Abstract:Besides solving the continuous optimization problems, this chapter introduces the evolutionary multitasking algorithm for solving the complex combinatorial optimization problems. In particular, in this chapter, we first present a generalized variant of vehicle routing problem with occasional drivers, i.e., Vehicle Routing Problem with Heterogeneous capacity, Time window and Occasional driver (VRPHTO), which is inspired by today’s “crowdshipping” and “sharing economy” in vehicle routing. Next, to further conceptualize the cloud-based optimization service that is capable of catering to multiple VRPHTOs requests at the same time, we present an evolutionary multitasking algorithm (EMA) to optimize multiple VRPHTOs simultaneously.

Abstract:Recently, evolutionary multitasking (EMT) has been proposed in the field of evolutionary computation as a new search paradigm, for solving multiple optimization tasks simultaneously. By sharing useful traits found along the evolutionary search process across different optimization tasks, the optimization performance on each task could be enhanced. The autoencoding-based EMT is a recently proposed EMT algorithm. In contrast to most existing EMT algorithms, which conduct knowledge transfer across tasks implicitly via crossover, it intends to perform knowledge transfer explicitly among tasks in the form of task solutions, which enables the employment of task-specific search mechanisms for different optimization tasks in EMT. However, the autoencoding-based explicit EMT can only work on continuous optimization problems. It will fail on combinatorial optimization problems, which widely exist in real-world applications, such as scheduling problem, routing problem, and assignment problem. To the best of our knowledge, there is no existing effort working on explicit EMT for combinatorial optimization problems. Taking this cue, in this article, we thus embark on a study toward explicit EMT for combinatorial optimization. In particular, by using vehicle routing as an illustrative combinatorial optimization problem, the proposed explicit EMT algorithm (EEMTA) mainly contains a weighted $l_{1}$ -norm-regularized learning process for capturing the transfer mapping, and a solution-based knowledge transfer process across vehicle routing problems (VRPs). To evaluate the efficacy of the proposed EEMTA, comprehensive empirical studies have been conducted with the commonly used vehicle routing benchmarks in multitasking environment, against both the state-of-the-art EMT algorithm and the traditional single-task e-olutionary solvers. Finally, a real-world combinatorial optimization application, that is, the package delivery problem (PDP), is also presented to further confirm the efficacy of the proposed algorithm.

Abstract:Multifactorial optimization (MFO) is a new paradigm proposed recently for evolutionary multi-tasking. In contrast to traditional evolutionary optimization approaches, which focus on solving only a single optimization problem at a time, MFO was proposed to solve multiple optimization problems simultaneously. It is contended that the concept of evolutionary multi-tasking provides the scope for implicit knowledge transfer of useful traits across different but related problem domains, thereby enhancing the evolutionary search for problem-solving. With the aim of evolutionary multi-tasking, multifactorial evolutionary algorithm (MFEA) was proposed in [1], and demonstrated efficient multi-tasking performances on several problem domains, including continuous, discrete, and the mixtures of continuous and combinatorial tasks. To solve different problems, the design of unified solution representations and effective problem specific decoding operators are required in MFEA. In particular, the random-key unified representation and the sorting based decoding operator were presented in MFEA for multi-tasking in the context of vehicle routing problem. However, problems such as ineffective solution representation and decoding are existed in this unified representation, which would deteriorate the multi-tasking performance of MFEA. Taking this cue, in this paper, we propose an improved MFEA (P-MFEA) with a permutation based unified representation and a split based decoding operator. To evaluate the efficacy of the proposed P-MFEA, comparison against the traditional single task evolutionary search paradigm on 12 multi-tasking capacitated vehicle routing problems is presented and discussed.

Abstract:Aiming at the Vehicle Scheduling Problem with non-full load,the paper has proposed a kind of adaptive genetic algorithm based on Grefenstette coding.This coding method can make any of genotype individual of operation correspondent to a travel route with real significance after crossover operator and mutation operation.During the crossover operator and mutation operation,premature convergence and destruction of chromosome are avoided by introducing self-adaptation adjust tactics.The simulation shows that the algorithm proposed in this paper is effective compared with simple genetic algorithm.
Matheuristic for a Two-Echelon Capacitated Vehicle Routing Problem with Environmental Considerations in City Logistics Service

Abstract:This paper addresses a two-echelon capacitated vehicle routing problem (2E-CVRP) with environmental considerations (2E-CVRP-E). A new arc-and-route-based mathematical model is constructed to formulate the problem in which the sum of drivers' wage, fuel cost, and handling cost is minimized. A matheuristic based on variable neighborhood search (VNS) and integer programming is designed to solve the 2E-CVRP-E. The integer programming in the matheuristic is used as a post-optimization technique to find better solutions missed by the VNS algorithm or to construct the least-cost first-level routes. To validate its effectiveness, the matheuristic first performs tests on 2E-CVRP instances and improves 13 current best-known solutions out of 234 instances. Then it performs tests on the 2E-CVRP-E instances modified from the 2E-CVRP. For 2E-CVRP-E instances, the total cost of the best solution found by the matheuristic is smaller than that of the best-known 2E-CVRP solution with an average relative gap of 6.37%. Computational results prove that the proposed matheuristic can find high-quality solutions for the 2E-CVRP and the 2E-CVRP-E.

Abstract:The capacitated vehicle routing problem studied in this paper stems from an e-commerce company in China. Efficient delivery is crucial for the logistic service of the company. It was observed that experienced drivers (experts) planned better delivery routes than those from optimization tools. This is largely due to the fact that the objectives (or the cost matrices) in real life are highly complicated and the experts use more practical objectives while making decisions. In this paper, we propose an inverse optimization formulation to derive a proper cost matrix by learning from the experts experience. Thus, the routing model with respect to the learned cost matrix could provide solutions as good as those given by experts. A multiplicative weights updates algorithm is applied to achieve a fast and convergent learning process. Experimental analyses based on randomly generated instances and real-world instances demonstrate the effectiveness of the approach. (c) 2021 Elsevier B.V. All rights reserved.

Abstract:With the emergence of crowdshipping and sharing economy, vehicle routing problem with occasional drivers (VRPOD) has been recently proposed to involve occasional drivers with private vehicles for the delivery of goods. In this article, we present a generalized variant of VRPOD, namely, the vehicle routing problem with heterogeneous capacity, time window, and occasional driver (VRPHTO), by taking the capacity heterogeneity and time window of vehicles into consideration. Furthermore, to meet the requirement in today's cloud computing service, wherein multiple optimization tasks may need to be solved at the same time, we propose a novel evolutionary multitasking algorithm (EMA) to optimize multiple VRPHTOs simultaneously with a single population. Finally, 56 new VRPHTO instances are generated based on the existing common vehicle routing benchmarks. Comprehensive empirical studies are conducted to illustrate the benefits of the new VRPHTOs and to verify the efficacy of the proposed EMA for multitasking against a state-of-art single task evolutionary solver. The obtained results showed that the employment of occasional drivers could significantly reduce the routing cost, and the proposed EMA is not only able to solve multiple VRPHTOs simultaneously but also can achieve enhanced optimization performance via the knowledge transfer between tasks along the evolutionary search process.

Abstract:In this chapter, a new dynamic capacitated arc routing problem (CARP) is defined and investigated. Compared with the static CARP and other dynamic CARP investigated by the existing researches, the new dynamic CARP is more general and closer to reality, and thus is more worthwhile to be solved. Due to the stochastic factors included in the dynamic CARP, the objective is not to obtain the optimal solution in a specific environment, but to find a robust solution that shows good performance in all the possible environments. For the dynamic CARP, a robustness measure based on repair operator is defined. The corresponding repair operator is designed according to the real-world considerations. Then, the benchmark instances of the dynamic CARP are generated by extending from the static counterparts to facilitate evaluating potential approaches. After that, the preliminary analysis for the fitness landscape of the dynamic CARP is conducted by experimental studies.

Abstract:The capacitated electric vehicle routing problem is a challenging non-deterministic polynomial hard (NP-hard) problem consisting of two interdependent sub-problems, the routing optimization problem and the charging decision problem. The routing optimization for electric vehicles with limited driving range is dependent on the available charging stations, while the charging decision is based on the charging demand that is estimated on the fixed route in return. Taking this coupling relationship into consideration, this paper proposes a dual-population based co-evolutionary algorithm that uses two evolution populations to collaboratively optimize these two sub-problems. In routing population, the charging station is regarded as a kind of customer with no demand, and an improved ant colony optimization algorithm is designed to generate routes that involve the position information of charging stations. In charging population, a binary genetic algorithm is used to generate a population of charging schemes whose qualities are evaluated based on the best ant obtained from the routing population, and then the resultant solution by inserting the best charging scheme is used to update the pheromone for the routing generation. Through the information interaction during the evolution, these two populations collaboratively search for the optimal solution of the problem. Experimental results demonstrate that the proposed algorithm can be able to avoid falling into the local optimum and has a reduction of about 4% in route distance averaged over two test suites. Additionally, it also has a high computational efficiency, which is faster than the advanced ant colony optimization method by about 2 times.

Abstract:The capacitated vehicle routing problem (CVRP) aims to find the routes that minimize transportation costs. However, in real-world applications, the equitable workload is essential for the drivers and logistics companies. For assigning an appropriate load for each vehicle, this paper formulates the CVRP with workload balancing as a multi-objective optimization problem (MO-CVRP). The goal is to simultaneously minimize the total length of routes and the variance of loads assigned to each vehicle. Although several multi-objective evolutionary algorithms (MOEAs) have been proposed for the MO-CVRP, they often suffer from slow convergence speeds due to the complexity of the search space, which hinders the identification of clear search directions. To address this issue, the knowledge transfer method is introduced that can leverage search experiences from related problems to expedite the solution process of the current problem. Specifically, a co-evolutionary genetic algorithm with knowledge transfer is proposed, where a simplified version of the traveling salesman problem (TSP) by disregarding the vehicle capacity constraint is utilized to facilitate the quick solution of the original MO-CVRP. To enable information interaction between these two problems, the widely used denoising autoencoder is adopted to construct a transformation relation between solutions from the TSP to the MO-CVRP. Additionally, an adaptive migration strategy is proposed to adaptively select the migration methods and an improved split operator strategy is designed to ensure the feasibility of the solutions. The proposed algorithm is compared with four state-of-the-art MOEAs on MO-CVRP test sets with different scales. Experimental results show that the proposed algorithm exhibits faster convergence speed and achieves solutions with superior convergence.

Abstract:A hybrid optimization algorithm is presented to solve capacitated vehicle routing problem. In the hybrid algorithm, chaotic particle swarm optimization (CPSO) adopts chaotic mapping and combines local search (by self experience) and global search (by neighboring experience) to search the optimal results and simulated annealing (SA) algorithm employs certain probability to avoid becoming trapped in a local optimum. The results obtained from the computational study show that the proposed algorithm is a feasible and effective method for capacitated vehicle routing problem.

Abstract:The capacitated arc routing problem (CARP) is a challenging vehicle routing problem with numerous real world applications. In this paper, an extended version of CARP, the multidepot capacitated arc routing problem (MCARP), is presented to tackle practical requirements. Existing CARP heuristics are extended to cope with MCARP and are integrated into a novel evolutionary framework: the initial population is constructed either by random generation, the extended random path-scanning heuristic, or the extended random Ulusoy's heuristic. Subsequently, multiple distinct operators are employed to perform selection, crossover, and mutation. Finally, the partial replacement procedure is implemented to maintain population diversity. The proposed evolutionary approach (EA) is primarily characterized by the exploitation of attributes found in near-optimal MCARP solutions that are obtained throughout the execution of the algorithm. Two techniques are employed toward this end: the performance information of an operator is applied to select from a range of operators for selection, crossover, and mutation. Furthermore, the arc assignment priority information is employed to determine promising positions along the genome for operations of crossover and mutation. The EA is evaluated on 107 instances with up to 140 nodes and 380 arcs. The experimental results suggest that the integrated evolutionary framework significantly outperforms these individual extended heuristics.

Abstract:The Capacitated Vehicle Routing Problem (CVRP) is a widely investigated NP-hard problem, which aims to determine the routes for a fleet of vehicles to serve a group of customers with minimum travel cost. In this paper, a fast evolutionary algorithm is proposed to solve CVRPs. To this end, a relevance matrix storing the probability that two customers are served successively by the same vehicle is calculated according to the local information of customer location and elite individuals in population. Based on the relevance matrix, an evolutionary algorithm called RMEA is proposed, where the relevance matrix is used to guide the crossover operation and accelerate the convergence of algorithm. Moreover, a relevance matrix based diversity preservation strategy is designed to increase the population diversity and solution quality. In the experiments, the proposed RMEA is compared to eight state-of-the-art heuristic methods tailored for CVRPs. Experimental results on three CVRP benchmarks demonstrate that the proposed RMEA is superior over eight compared algorithms and shows fast convergence speed.

Abstract:The Internet of Things integrates lots of capacitated vehicles in smart logistics. The routing for capacitated vehicles is a combinatorial optimization problem which has been widely studied in recent years. This paper proposes an effective order-aware hybrid genetic algorithm for the capacitated vehicle routing problem in the Internet of Things. The method is characterized by an improved initialization strategy and a problem-specific crossover operator. The former combines the sweep algorithm with randomness to harmonize the contradiction between diversity and convergence, while the latter integrates neighborhood search heuristics to find the offspring with the best fitness and check constraints simultaneously. A large number of simulations have been carried out, and the results validated the effectiveness of our algorithm.

Abstract:The cumulative capacitated vehicle routing problem with single (CCVRP) or multiple depots (MDCCVRP) is a variant of the popular capacitated vehicle routing problem. Instead of minimizing the total travel time, the objective here is to minimize the sum of all customers’ waiting times. This problem has a variety of real-world applications, especially in post-disaster humanitarian relief. To solve the challenging CCVRP and MDCCVRP, we propose a unified two-individual evolutionary algorithm that follows the memetic search framework. The algorithm integrates several key features: a two-individual population mechanism to accelerate convergence while maintaining population diversity, a dedicated edge assembly crossover to generate high-quality offspring and an adaptive feasible and infeasible local search to achieve a balanced exploration between feasible and infeasible solutions. The algorithm is evaluated on 39 CCVRP instances and 78 MDCCVRP instances commonly used in the literature. Computational results show that for the CCVRP, the algorithm outperforms the leading algorithms by achieving improved best results (new upper bound) for 13 instances and matching the best results for 23 other instances. For the MDCCVRP, the algorithm achieves 9 improved best results and matches the best results for the remaining instances. The critical components of the algorithm are investigated to understand their contributions.

A two-level algorithm for capacitated vehicle routing problem with three-dimensional loading constraints

Abstract:This paper addresses a variation of the capacitated vehicle routing problem, known as the Capacitated Vehicle Routing Problem with Three-Dimensional Loading Constraints (3L-CVRP), which is a highly complex combinatorial optimization problem. We solve this problem with a two-level algorithm, consisting of an outer stage and an inner stage. A tabu search algorithm is developed for the outer stage which handles the vehicle routing problem, whereas a loading check algorithm for searching the residual capacity of a vehicle is developed for the inner stage. We consider a new space structure based on the support area for the design of the loading check algorithm. The space structure, coupled with three loading strategies, provides more options for handling different loading scenarios. The proposed algorithm is tested by solving some benchmark instances and yields results that are better on average than the existing best solutions obtained from other approaches.

Abstract:Vehicle routing problem (VRP) is a well-known NP-hard combinational optimization problem. In the literature, existing approaches can be generally classified into two categories: exact methods and metaheuristics methods. The former is only effective for small problem instances while the latter is more suitable for practical applications with larger scale. However, these methods perform evolutionary search only on a single problem form of VRP, while the efficient problem form of a given VRP is often unknown before hand. Keeping the above in mind, this paper proposes memetic search with evolutionary multitasking for solving vehicle routing problem on multiple problem forms. In particular, multiple simplified vehicle routing problems are firstly constructed and acted as the auxiliary tasks of original VRP. The memetic evolutionary search is thus simultaneously performed on simplified vehicle routing problems and original VRP. In this way, the useful routing traits can be shared by knowledge transfer among the tasks to enhance the evolutionary search. To verify the performance of the proposed method, comprehensive empirical experiments have been conducted on commonly used VRP benchmarks.
