Abstract:Target detection is one of the most important applications in hyperspectral remote sensing image analysis. Sparse representation method has been considered to be effective in hyperspectral target detection. In this method, a sparse representation with respect to a certain pixel in hyperspectral imagery means a linear combination of few data vectors in the data dictionary. An training dictionary consisting of both target and background samples in the same feature space is first constructed and test pixels are sparsely represented by decomposing over the dictionary. Though sparse representation is considered to preserve main information of most pixels, inevitable indeterminacy may lead to different representations of same or similar pixels. In this paper, a manifold regularized sparsity model is proposed to deal with this problem. A graph regularization term is incorporated into the sparsity model under the manifold assumption that similar data pixels should have similar sparse representation. Then a modified simultaneous version of the SP algorithm (SSP) is implemented to obtain the recovered sparse vectors which are composed of sparse coefficients corresponding to both target sub-dictionary and background sub-dictionary. Once the sparse vectors are obtained, the residual between original test samples and estimate recovered from target sub-dictionary as well as the residual between original test samples and estimate recovered from background sub-dictionary are calculated to determine the test pixels' class. The proposed algorithm is applied to real hyperspectral image to detect targets of interest. Experimental results show a more accurate target detection performance with this proposed model over that with conventional sparse models.

Abstract:Target detection is a crucial problem for the analysis of hyperspectral remote sensing image. Sparse representation-based methods have shown considerable potential in hyperspectral target detection. In a hyperspectral image (HSI), the sparse representation with respect to a certain pixel means the pixel can be sparsely represented by the linear combination of data vectors from the data dictionary. When applied to target detection, a training dictionary needs to be constructed, consisting of both target and background samples in the same feature space. Then the test pixels can be sparsely represented through the decomposition over the constructed dictionary. Sparse representation is considered to preserve the main information of most pixels in HSI target detection. However, some background pixels may possess spectra similar to the target pixels' spectra, which may cause false detection. Therefore, more constraints are needed to smooth these pixels. We propose a local similarity constraint-based sparse algorithm to deal with this problem. Based on the assumption that pixels have both spectral and spatial similarity should have similar sparse representation, a local similarity constraint term is incorporated into the sparsity model. Then, an iterative sparse recovery algorithm is provided to obtain the recovered sparse vectors composed of sparse coefficients corresponding to both the target subdictionary and the background subdictionary. With the obtained sparse vectors, the residuals between the original test samples and the estimates recovered from the dictionary (including the target subdictionary and the background subdictionary) can be calculated and used to decide which class the test pixels belong to. The proposed algorithm has been applied on real HSIs to test the performance of detecting targets of interest. Experimental results demonstrate that the proposed model achieves better target detection performance than the state-of-the-art methods. Attention-based Sparse and Collaborative Spectral Abundance Learning for Hyperspectral Subpixel Target Detection

Abstract:The subpixel target detection in hyperspectral image processing persists as a formidable challenge. In this paper, we present a novel subpixel target detector termed attention-based sparse and collaborative spectral abundance learning for subpixel target detection in hyperspectral images. To help suppress background during subpixel target detection, the proposed method presents a pixel attention-based background sample selection method for background dictionary construction. Besides, the proposed method integrates a band attention-based spectral abundance learning model, replete with sparse and collaborative constraints, in which the band attention map can contribute to enhancing the discriminative ability of the detector in identifying targets from backgrounds. Ultimately, the detection result of the proposed detector is achieved by the learned target spectral abundance after solving the designed model using the alternating direction method of multipliers algorithm. Rigorous experiments conducted on four benchmark datasets, including one simulated and three real-world datasets, validate the effectiveness of the detector with the probability of detection of 90.88%, 96.86%, and 97.79% on the PHI, RIT Campus, and Reno Urban data, respectively, under fixed false alarm rate equal 0.01, indicating that the proposed method yields superior hyperspectral subpixel detection performance and outperforms existing methodologies.

Abstract:Hyperspectral images provide great potential for target detection, however, new challenges are also introduced for hyperspectral target detection, resulting that hyperspectral target detection should be treated as a new problem and modeled differently. Many classical detectors are proposed based on the linear mixing model and the sparsity model. However, the former type of model cannot deal well with spectral variability in limited endmembers, and the latter type of model usually treats the target detection as a simple classification problem and pays less attention to the low target probability. In this case, can we find an efficient way to utilize both the high-dimension features behind hyperspectral images and the limited target information to extract small targets? This paper proposes a novel sparsity-based detector named the hybrid sparsity and statistics detector (HSSD) for target detection in hyperspectral imagery, which can effectively deal with the above two problems. The proposed algorithm designs a hypothesis-specific dictionary based on the prior hypotheses for the test pixel, which can avoid the imbalanced number of training samples for a class-specific dictionary. Then, a purification process is employed for the background training samples in order to construct an effective competition between the two hypotheses. Next, a sparse representation-based binary hypothesis model merged with additive Gaussian noise is proposed to represent the image. Finally, a generalized likelihood ratio test is performed to obtain a more robust detection decision than the reconstruction residual-based detection methods. Extensive experimental results with three hyperspectral data sets confirm that the proposed HSSD algorithm clearly outperforms the state-of-the-art target detectors.

Abstract:<p>The performance of subspace-based methods such as matched subspace detector (MSD) and MSD with interaction effects (MSDinter) heavily depends on the background subspace and the target subspace. Nonetheless, constructing a representative target subspace is challenging due to the limited availability of target spectra in a collected hyperspectral image. In this paper, we propose two new hyperspectral target detection methods termed data-augmented MSD (DAMSD) and data-augmented MSDinter (DAMSDI) that can effectively solve the scarcity problem of target spectra and from which a representative target-background mixed subspace can be learned. We first synthesise target-background mixed spectra based on classical hyperspectral mixing models and then learn a target-background mixed subspace via principal component analysis. Compared with MSD and MSDinter, the learned mixed subspace is more representative as spectral variability of target spectra is explained to the largest extent and it leads to an improvement in computational speed and numerical stability. We demonstrate the efficacy of DAMSD and DAMSDI for subpixel target detection on two public hyperspectral image datasets.</p>

Abstract:Due to the limitations of hardware technology and budget constraints, there always exists a tradeoff between spatial and spectral resolutions in a hyperspectral image (HSI). Because of the limited spatial resolution, mixed pixels are a common issue in HSIs, and consequently, some targets appear as subpixels. The effectiveness of hyperspectral target detection is affected greatly by the subpixel targets, especially when the size of the targets is small. In this article, we proposed a double dictionary-based nonlinear representation model for hyperspectral subpixel target detection (DDNRTD). DDNRTD represents HSIs with a nonlinear model based on background and target dictionaries, which fully considers the spatial property of background and targets and can separate background and targets reliably, especially for small-sized subpixel targets. In addition, we designed an over-completed background dictionary construction strategy to represent the background part more effectively, which integrates spectral angle distance (SAD) with sparse representation. Experiments on two simulated and five real HSI datasets showed that the proposed DDNRTD method produced more accurate detection results than six state-of-the-art methods.

Hyperspectral Anomaly Detection with Data Sphering and Unsupervised Target Detection.

Abstract:Low rank and sparse representation (LRaSR)-based approaches have been widely used for hyperspectral anomaly detection (HAD) by effectively decomposing a hyperspectral data set into a low - rank component for background (BKG), a sparse component for anomalies, and a residual component for noise. This paper proposed a novel hyperspectral anomaly detection (AD) method based on data sphering (DS) and unsupervised target detection with sparse cardinality (DS-UTSSC). First of all, DS-UTS uses data sphering to remove BKG, which is characterized by 1 st and 2 nd statistics, for original data $X$ . Second, potential anomaly component $\mathrm{S}_{\text{DS}-\mathrm{U}\text{TS}}$ is generated via unsupervised target detection and subspace projection for the sphered data $X$ . To further reduce the impact of noise on anomaly detection, sparse cardinality (SC) is incorporated to obtain $\mathrm{S}_{\text{DS}-\text{UTSSC}}$ . Finally, RX-AD is implemented on $\mathrm{S}_{\mathrm{D}\text{S-UTSSC}}$ to detect anomalies. The experimental results validate that DS-UTSSC is very competitive against the LRaSR-based models and AE-based method.
Linear Feature Detection for Hyperspectral Subpixel Mapping

Abstract:The ignorance of the spatial structure of subpixel is one of the factors that influence the accuracy of hyperspectral subpixel mapping. In order to effectively solve this problem, a subpixel mapping algorithm is proposed that based on linear feature detection in mixed pixels. Firstly, the mixed pixels of typical linear feature classes are determined by spectral unmixing. Then, based on the maximum linear index method of the complete straight-line set, the linear features of remaining mixed pixels are determined. The template matching method is used in conjunction with the pixel attraction to determine the classes of linear subpixels. Finally, the subpixel categories of the remaining mixed pixels are iteratively determined based on the linear optimization method. The experimental results of real data and simulation data show that the proposed method can effectively improve the precision of subpixel mapping.

Abstract:Recent studies indicate sparse representation has achieved very good results in hyperspectral imaging tar-get detections. However, sparse representation only uses the spectral information of the hyperspectral imaging, with-out considering the spatial information. The purpose of this paper is to research the influence of hyperspectral ima-ging's spatial correlation on the target detection algorithm, and propose two new sparse representation models, which named 4-neighborhood smoothing sparse model and 4-neighborhood union sparse model, considering sparse representation of both target pixels and its 4-neighborhood pixels to improve the effectiveness and efficiency of the target detection algorithm. With three real hyperspectral imaging datasets in the simulation experiment, the results show that the algorithms utilizing the new models could improve the effectiveness or efficiency of the test results to a certain degree.

Abstract:A kernel-based signature space orthogonal projection(KSSP) technique is proposed for nonlinear subpixel target detection in hyperspectral imagery.As a nonlinear version of the signature space orthogonal projection(SSP),the SSP is adopted in a high-dimension feature space after the pixels of input space are mapped into the feature space via nonlinear mapping.The kernel trick allows the KSSP ignor the actual nonlinear mapping.Experimental results of simulated and real data prove that the proposed KSSP approach outperforms the SSP method in target detection,and improves the robustness to noise.

Abstract:The high dimensionality of a hyperspectral image (HSI) provides the possibility of deeply capturing the underlying and intrinsic characteristics in spectra, such that targets embedded in the background can be detected. However, redundant information, deteriorated bands, and other interferences from background challenge the target detection problem. In this article, an effective feature extraction method based on unsupervised networks is proposed to mine intrinsic properties underlying HSIs. Our approach, called spectral regularized unsupervised networks (SRUN), imposes spectral regularization on autoencoder (AE) and variational AE (VAE) to emphasize spectral consistency, which is more suitable for characterizing spectral information of HSIs by hidden nodes than the original AE and VAE models. Then, we conduct a simple feature selection algorithm on the hidden nodes in the deepest code to select specific nodes that contain distinguishability between target and background, which is based on the spectral angular difference between a known target spectrum and spectra of other pixels in input. The selected nodes are further weighted adaptively to obtain a discriminative map depending on the observation that each selected node provides different contribution rates to target detection. Experimental results on several data sets illustrate that the proposed SRUN-based target detection algorithm is suitable for targets at the subpixel level and those with structural information.

Abstract:Abundant spectral information endows unique advantages of hyperspectral remote sensing images in target location and recognition. Target detection techniques locate materials or objects of interest from hyperspectral images with given prior target spectra, and have been widely used in military, mineral exploration, ecological protection, etc. However, hyperspectral target detection is a challenging task due to high-dimension data, spectral changes, spectral mixing, and so on. To this end, many methods based on optimization and machine learning have been proposed in the past decades. In this paper, we review the representatives of hyperspectral image target detection methods and group them into seven categories: hypothesis testing-based methods, spectral angle-based methods, signal decomposition-based methods, constrained energy minimization (CEM)-based methods, kernel-based methods, sparse representation-based methods, and deep learning-based methods. We then comprehensively summarize their basic principles, classical algorithms, advantages, limitations, and connections. Meanwhile, we give critical comparisons of the methods on the summarized datasets and evaluation metrics. Furthermore, the future challenges and directions in the area are analyzed.

Hyperspectral Target Detection Based on Tensor Sparse Representation

Abstract:The sparse representation-based detection (SRD) algorithm has already shown the effectiveness for hyperspectral target detection (TD) recently. However, SRD does not utilize spatial information of hyperspectral imagery (HSI). In this letter, a novel tensor SRD (TSRD) algorithm is proposed to take jointly the spatial and the spectral information of HSI into account. TSRD extends each atom of both the target and the background dictionaries into a third-order tensor where the local spatial neighborhood information can be well preserved. It not only possesses the advantages of SRD that no assumptions about the target and background distributions are required and spectral variability can be considered but also exploits the spatial information of HSI to further increase the accuracy of TD. The experimental results on both synthetic and real hyperspectral data show that the proposed TSRD method outperforms traditional and state-of-the-art TD methods in terms of detection accuracy.
Composite Kernel Target Detection Based on Mathematical Morphology for Hyperspectral Imagery

Abstract:In the base of kernel signature space orthogonal projection (KSSP), a composite kernel signature space orthogonal projection (CKSSP) technique, which combines spectral information with spatial information, is proposed for target detection in nonlinearly mixed hyperspectral imagery. The grey mathematical morphological transform is extended into multivariate mathematical morphological transform based on marginal ordering and reduced ordering, respectively. The pixel distance is used as ordering scale function to establish reduced ordering. Extended mathematical morphological method with multi-structure elements is used to extract spatial information of hyperspectral images. Combining the spectral and spatial information, the composite kernel function is constructed and improved according to kernel function definition. Target is detected by CKSSP. The proposed method not only sufficiently applies the spectral information, but also effectively takes into account the spatial information. Experimental results of simulated data demonstrate that root mean square error of CKSSP is 0.03 less than that of KSSP, Experimental results of real data and the receiver operating characteristic curves show that CKSSP approach slightly outperforms the KSSP method in target detection.
Self-supervised spectral matching network for hyperspectral target detection

Abstract:Hyperspectral target detection is a pixel-level recognition problem. Given a few target samples, it aims to identify the specific target pixels such as airplane, vehicle, ship, from the entire hyperspectral image. In general, the background pixels take the majority of the image and complexly distributed. As a result, the datasets are weak annotated and extremely imbalanced. To address these problems, a spectral mixing based self-supervised paradigm is designed for hyperspectral data to obtain an effective feature representation. The model adopts a spectral similarity based matching network framework. In order to learn more discriminative features, a pair-based loss is adopted to minimize the distance between target pixels while maximizing the distances between target and background. Furthermore, through a background separated step, the complex unlabeled spectra are downsampled into different sub-categories. The experimental results on three real hyperspectral datasets demonstrate that the proposed framework achieves better results compared with the existing detectors.

Abstract:The detection and identification of target pixels such as certain minerals and man-made objects from hyperspectral remote sensing images is of great interest for both civilian and military applications. However, due to the restriction in the spatial resolution of most airborne or satellite hyperspectral sensors, the targets often appear as subpixels in the hyperspectral image (HSI). The observed spectral feature of the desired target pixel (positive sample) is therefore a mixed signature of the reference target spectrum and the background pixels spectra (negative samples), which belong to various land cover classes. In this paper, we propose a novel supervised metric learning (SML) algorithm, which can effectively learn a distance metric for hyperspectral target detection, by which target pixels are easily detected in positive space while the background pixels are pushed into negative space as far as possible. The proposed SML algorithm first maximizes the distance between the positive and negative samples by an objective function of the supervised distance maximization. Then, by considering the variety of the background spectral features, we put a similarity propagation constraint into the SML to simultaneously link the target pixels with positive samples, as well as the background pixels with negative samples, which helps to reject false alarms in the target detection. Finally, a manifold smoothness regularization is imposed on the positive samples to preserve their local geometry in the obtained metric. Based on the public data sets of mineral detection in an Airborne Visible/Infrared Imaging Spectrometer image and fabric and vehicle detection in a Hyperspectral Mapper image, quantitative comparisons of several HSI target detection methods, as well as some state-of-the-art metric learning algorithms, were performed. All the experimental results demonstrate the effectiveness of the proposed SML algorithm for hyperspectral target detection.

Abstract:The Multiple Instance Hybrid Estimator for discriminative target characterization from imprecisely labeled hyperspectral data is presented. In many hyperspectral target detection problems, acquiring accurately labeled training data is difficult. Furthermore, each pixel containing target is likely to be a mixture of both target and non-target signatures (i.e., sub-pixel targets), making extracting a pure prototype signature for the target class from the data extremely difficult. The proposed approach addresses these problems by introducing a data mixing model and optimizing the response of the hybrid sub-pixel detector within a multiple instance learning framework. The proposed approach iterates between estimating a set of discriminative target and non-target signatures and solving a sparse unmixing problem. After learning target signatures, a signature based detector can then be applied on test data. Both simulated and real hyperspectral target detection experiments show the proposed algorithm is effective at learning discriminative target signatures and achieves superior performance over state-of-the-art comparison algorithms.

Abstract:Hyperspectral images (HSIs) can provide discriminative spectral signatures regarding the physical nature of different materials. It is this unique nature that makes HSIs to be of great interest in many fields. However, HSI application faces various challenges due to high dimensionality, redundant information, noisy bands, and insufficient samples. To address these problems, we propose an unsupervised band selection method based on deep latent spectral representation learning, called DLSRL, in this article. It imposes spectral consistency on deep latent space that resolves the issue of insufficient samples and spectral information lost in HSI interpretation. It pursues the low-dimensional optimal representation of the high-dimensional HSIs. In particular, an adaptive mapping relationship is constructed between the deep latent representation and the optimal subset to preserve physical significance optimally. Furthermore, a hierarchical optimization approach is introduced to achieve target detection with the selected subset. To verify the superiority of the proposed method, experiments have been conducted on four data sets captured by different sensors over different scenes. Comparative analyses validate that the proposed method presents superior performance in terms of high detection accuracy and low false alarm rate.

Abstract:In recent years, with the development of compressed sensing theory, sparse representation methods have been concerned by many researchers. Sparse representation can approximate the original image information with less space storage. Sparse representation has been investigated for hyperspectral imagery (HSI) detection, where approximation of testing pixel can be obtained by solving l1-norm minimization. However, l1-norm minimization does not always yield a sufficiently sparse solution when a dictionary is not large enough or atoms present a certain level of coherence. Comparatively, non-convex minimization problems, such as the lp penalties, need much weaker incoherence constraint conditions and may achieve more accurate approximation. Hence, we propose a novel detection algorithm utilizing sparse representation with lp-norm and propose adaptive iterated shrinkage thresholding method (AISTM) for lp-norm non-convex sparse coding. Target detection is implemented by representation of the all pixels employing homogeneous target dictionary (HTD), and the output is generated according to the representation residual. Experimental results for four real hyperspectral datasets show that the detection performance of the proposed method is improved by about 10% to 30% than methods mentioned in the paper, such as matched filter (MF), sparse and low-rank matrix decomposition (SLMD), adaptive cosine estimation (ACE), constrained energy minimization (CEM), one-class support vector machine (OC-SVM), the original sparse representation detector with l1-norm, and combined sparse and collaborative representation (CSCR).

Abstract:Owing to significantly improved spectral resolution, a hyperspectral imaging sensor can now uncover many unknown subtle material substances. In many cases, anomalies are usually embedded in the background. To develop a means through which these anomalies may be detected and separated from the background, we propose a spectral-spatial anomaly detection method based on a selected band subset. To be specific, we constrain an unsupervised network by making full use of the underlying physical characteristics which are beneficial to hyperspectral anomaly detection. Based on that, a selection criterion is constructed to adaptively select a subset of bands that essentially contain discriminative and informative features between the anomaly and background in an unsupervised manner. Then, the selected bands are simultaneously inputted into the spatial detector and spectral detector. To overcome the deficiencies of detecting anomalies in only one aspect, an adaptive combination of spatial result and the spectral result is introduced. Finally, a simple and powerful iterative suppression is conducted on the initial detection map to further reduce false alarm rate while ensuring detection capability. Extensive empirical researches performed on eighteen publicly available hyperspectral images (HSIs) of different sizes over different scenes demonstrate that our proposed method can achieve an average detection capability of 0.99564, and the average false alarm rate is one order of magnitude lower than the second one.
