Abstract:Community detection algorithms play an important role in revealing and analyzing complex network structures. However, when these algorithms are put into practice, privacy concerns often arise, especially when community nodes wish to safeguard their identities from exposure. This interaction between network analysis and privacy issues leads to what we refer to as the "community hiding problem." In the context of concealing specific target communities, popular methods primarily focus on preventing community detection algorithms from accurately identifying the entire original community, resulting in partial concealment. This study formally addresses the challenge of achieving complete concealment of target communities. We introduce key metrics such as escape scores, dispersion scores, and hiding scores to precisely define the problem. Additionally, we design a metric, denoted as M-value, to evaluate the effectiveness of concealing target communities from multiple perspectives. To tackle this challenge, we employ a genetic algorithm that leverages previous knowledge to maximize the concealment of the target community while minimizing changes to link connections. We validate our approach through extensive experiments with various real-world datasets, demonstrating that our algorithm outperforms several state-of-the-art baseline algorithms across multiple metrics. Visual representations of our method confirm its ability to effectively hide target communities while minimally affecting the broader network's community structure, strengthening the inherent effectiveness of our community hiding approach. Furthermore, we assess the adaptability of our modified network with different community detection algorithms, consistently demonstrating effective concealment even when these algorithms are extended. This emphasizes the robustness and generality of our proposed approach in various algorithmic scenarios.
Overlapping Community Hiding Method Based on Multi-Level Neighborhood Information

Abstract:The overlapping community detection algorithm divides social networks into multiple overlapping parts, and members can belong to multiple communities at the same time. Although the overlapping community detection algorithm can help people understand network topology, it exposes personal privacy. The BIH algorithm is proposed to solve the problem of personal privacy leaks in overlapping areas. However, some specific members in overlapping areas do not want to be discovered to belong to some specific community. To solve this problem, an overlapping community hiding algorithm based on multi level neighborhood information (MLNI) is proposed. The MLNI algorithm defines node probability of community based on multi-layer neighborhood information. By adjusting the probability of the target node belonging to each community, the difference between the probability that the target node belongs to outside and inside the target community is maximized. This process can be regarded as an optimization problem. In addition, the MLNI algorithm uses the genetic algorithm to find the optimal solution, and finally achieves the purpose of moving the target node in the overlapping area out of a specific community. The effectiveness of the MLNI algorithm is demonstrated through extensive experiments and baseline algorithms. The MLNI algorithm effectively realizes the protection of personal privacy in social networks.
A unified framework of community hiding using symmetric nonnegative matrix factorization

Abstract:Community detection can help us to deeply understand community structures and reveal potential social relationships among members. However, as people's concerns over the excessive mining of personal information have grown, the idea of community hiding has been proposed for privacy protection. Most existing community hiding methods based on heuristic approaches and genetic algorithms ignore the generative process of the network and cannot provide a better explanation of the rationality of the hiding mechanism. In addition, they are not simultaneously applicable to the global community, target community, or target nodes. In this study, we address the community hiding problem on three scales: global community hiding (macroscopic), target community hiding (mesoscopic), and target node hiding (microscopic). We propose a unified community hiding framework (CH-SNMF) that can be applied to all three scales. The basic idea is to use symmetric nonnegative matrix factorization to describe the network generative mechanism. It has a potential clustering capability that can mine key links and link sets during the network generation process. Therefore, they can be used to disrupt community structures with minimal perturbation budgets. The experimental results show that CH-SNMF outperforms many advanced baseline methods and effectively protects organizational and individual privacy.

Abstract:In recent years, overlapping community detection algorithms have been paid more and more attention, which not only reveal the real social relations, but also expose the possible communication channels between communities. Those individuals (or people) in the overlapping area are very important to the communities that can promote communication between two or more communities. On the other hand, from the privacy perspective, some people may not want to be found out in the overlapping areas. With this in mind, we raise a question “Can individuals modify their relationships to avoid the community discovery algorithms locating them into overlapping areas?” If this problem could be solved, these people may not need to worry about being disturbed. In particular, we first give three heuristic hiding strategies, i.e., Random Hiding(RH), Based Degree Hiding(DH) and Betweenness Hiding(BH), as comparison, utilizing the randomly the node, information of node degree and node betweenness centrality, respectively. And then, we propose a novel hiding algorithm by exploiting the importance degree of nodes in communities based on which the corresponding social connections are added or deleted called name BIH . Through extensive experiments, we show the effectiveness of the proposed algorithm in moving out a target node from overlapped areas.

Abstract:Community detection can reveal real social relations and enable great economic benefits for enterprises and organizations; however, it can also cause privacy problems such as the disclosure of individual or group information amongst community members, which goes against the hidden wishes of individuals and groups. Therefore, community hiding has received increasingly more attention in recent years. However, the network generation mechanism has not been considered in previous studies on community hiding. Generation models can reflect the generation process of the network and show the strength of the connection between nodes. To this end, we propose a new graph autoencoder for the community hiding algorithm, namely, GCH, which not only hides the community structure but also embodies the generation mechanism of the network. It uses the rules of the generation process from underfitting to overfitting in the community network to select the connections that have the greatest impact on the community structure for rewiring. After analyzing the essence of community detection algorithms and graph neural networks, an improved graph autoencoder is used to reconstruct the probabilistic adjacency matrix; and under the constraint of an ”invisible perturbation” of the network structure, the existing mainstream community detection algorithm is attacked, which greatly reduces the accuracy of community detection results. For the verification of model effectiveness, two widely used indicators NMI and AE are used to compare the performance of our attack on the community detection algorithm with other baselines under different dimension settings. Compared with several baseline algorithms, extensive experimental results are obtained.

Abstract:In the context of big data, user data have been released on the Internet on a large scale. Although these data always adopt anonymous ID, the corresponding user's real identification and other private information are still exposed to possible violations by attackers with certain background knowledge. In order to protect user's privacy, Samarita and Sweeny proposed k-anonymity model, which has been widely used in privacy protection. This model is mainly used in point-anonymization at this stage, and there is no good way for line-anonymization. This paper describes a method of anonymization based on genetic algorithm to protect the privacy of user's behavior pattern in stock BBS, which is a development of line-anonymization. Experimental results show that, the method described in this paper performs well in protecting privacy using k-anonymity model and has a controllable information loss.
Efficient Personalized Community Detection via Genetic Evolution

Abstract:Personalized community detection aims to generate communities associated with user need on graphs, which benefits many downstream tasks such as node recommendation and link prediction for users, etc. It is of great importance but lack of enough attention in previous studies which are on topics of user-independent, semi-supervised, or top-K user-centric community detection. Meanwhile, most of their models are time consuming due to the complex graph structure. Different from these topics, personalized community detection requires to provide higher-resolution partition on nodes that are more relevant to user need while coarser manner partition on the remaining less relevant nodes. In this paper, to solve this task in an efficient way, we propose a genetic model including an offline and an online step. In the offline step, the user-independent community structure is encoded as a binary tree. And subsequently an online genetic pruning step is applied to partition the tree into communities. To accelerate the speed, we also deploy a distributed version of our model to run under parallel environment. Extensive experiments on multiple datasets show that our model outperforms the state-of-arts with significantly reduced running time.

Abstract:Community detection plays an important role in social networks, since it can help to naturally divide the network into smaller parts so as to simplify network analysis. However, on the other hand, it arises the concern that individual information may be overmined, and the concept community deception has been proposed to protect individual privacy on social networks. Here, we introduce and formalize the problem of community detection attack and develop efficient strategies to attack community detection algorithms by rewiring a small number of connections, leading to privacy protection. In particular, we first give two heuristic attack strategies, i.e., Community Detection Attack (CDA) and Degree Based Attack (DBA), as baselines, utilizing the information of detected community structure and node degree, respectively. Then, we propose an attack strategy called "genetic algorithm (GA)-based Q-Attack," where the modularity Q is used to design the fitness function. We launch community detection attack based on the above three strategies against six community detection algorithms on several social networks. By comparison, our Q-Attack method achieves much better attack effects than CDA and DBA, in terms of the larger reduction of both modularity Q and normalized mutual information (NMI). In addition, we further take transferability tests and find that adversarial networks obtained by Q-Attack on a specific community detection algorithm also show considerable attack effects while generalized to other algorithms.

Abstract:Community structures contain important information of social networks. In most applications, mining community structures would be helpful for people to analyze networks. Typically, genetic algorithm is an effective approach to detect communities. At present, there are two kinds of genetic encoding methods: SGR (Tasgin et al., 2008) and LAR (Pizzuti, 2008) and both have some shortages, which always lead to premature convergence. Based on this, we proposed a new matrix encoding method for community detection, which contains total information of community clustering. We also designed crossover and mutation operator. Abstract:As the number of social network users grows exponentially with increasingly complex profiles, community detection algorithms play a critical role in user portrait analysis. The associated privacy concerns, however, have not sufficiently received the attention that it deserves. In this work, we investigate methods for obfuscating the original community structure by modifying a small number of connections imperceptibly so as to protect the privacy of users. The existing evolutionary models have some successes in this type of NP-hard problem but can only be applied to small-scale datasets, rendering them inadequate for real-world applications. To alleviate this problem, we propose an original and novel CoeCo, a cooperative evolutionary community obfuscation model. In CoeCo, we leverage the divide-and-conquer strategy and put forward a co-evolutionary optimization algorithm suitable for community structure, in which two different fitness functions promote each other to find the optimal edge set. In addition, the motif hypergraph and permanence are used to improve population initialization. The experimental results indicate that our proposed method can achieve excellent efficacy in obfuscating community structure and also greatly reduces running time.

Mechanisms for Hiding Sensitive Genotypes with Information-Theoretic Privacy

Abstract:Motivated by the growing availability of personal genomics services, we study an information-theoretic privacy problem that arises when sharing genomic data: a user wants to share his or her genome sequence while keeping the genotypes at certain positions hidden, which could otherwise reveal critical health-related information. A straightforward solution of erasing (masking) the chosen genotypes does not ensure privacy, because the correlation between nearby positions can leak the masked genotypes. We introduce an erasure-based privacy mechanism with perfect information-theoretic privacy, whereby the released sequence is statistically independent of the sensitive genotypes. Our mechanism can be interpreted as a locally-optimal greedy algorithm for a given processing order of sequence positions, where utility is measured by the number of positions released without erasure. We show that finding an optimal order is NP-hard in general and provide an upper bound on the optimal utility. For sequences from hidden Markov models, a standard modeling approach in genetics, we propose an efficient algorithmic implementation of our mechanism with complexity polynomial in sequence length. Moreover, we illustrate the robustness of the mechanism by bounding the privacy leakage from erroneous prior distributions. Our work is a step towards more rigorous control of privacy in genomic data sharing.
Evading Community Detection via Counterfactual Neighborhood Search

Abstract:Community detection techniques are useful for social media platforms to discover tightly connected groups of users who share common interests. However, this functionality often comes at the expense of potentially exposing individuals to privacy breaches by inadvertently revealing their tastes or preferences. Therefore, some users may wish to preserve their anonymity and opt out of community detection for various reasons, such as affiliation with political or religious organizations, without leaving the platform. In this study, we address the challenge of community membership hiding, which involves strategically altering the structural properties of a network graph to prevent one or more nodes from being identified by a given community detection algorithm. We tackle this problem by formulating it as a constrained counterfactual graph objective, and we solve it via deep reinforcement learning. Extensive experiments demonstrate that our method outperforms existing baselines, striking the best balance between accuracy and cost.

Abstract:Motivation: Researchers need a rich trove of genomic datasets that they can leverage to gain a better understanding of the genetic basis of the human genome and identify associations between phenotypes and specific parts of DNA. However, sharing genomic datasets that include sensitive genetic or medical information of individuals can lead to serious privacy-related consequences if data lands in the wrong hands. Restricting access to genomic datasets is one solution, but this greatly reduces their usefulness for research purposes. To allow sharing of genomic datasets while addressing these privacy concerns, several studies propose privacy-preserving mechanisms for data sharing. Differential privacy (DP) is one of such mechanisms that formalize rigorous mathematical foundations to provide privacy guarantees while sharing aggregated statistical information about a dataset. However, it has been shown that the original privacy guarantees of DP-based solutions degrade when there are dependent tuples in the dataset, which is a common scenario for genomic datasets (due to the existence of family members). Results: In this work, we introduce a near-optimal mechanism to mitigate the vulnerabilities of the inference attacks on differentially private query results from genomic datasets including dependent tuples. We propose a utility-maximizing and privacy-preserving approach for sharing statistics by hiding selective SNPs of the family members as they participate in a genomic dataset. By evaluating our mechanism on a real-world genomic dataset, we empirically demonstrate that our proposed mechanism can achieve up to 40% better privacy than state-of-the-art DP-based solutions, while near-optimally minimizing the utility loss.

Abstract:A social network is a platform that users can share data through the internet. With the ever-increasing intertwining of social networks and daily existence, the accumulation of personal privacy information is steadily mounting. However, the exposure of such data could lead to disastrous consequences. To mitigate this problem, an anonymous group structure algorithm based on community structure is proposed in this article. At first, a privacy protection scheme model is designed, which can be adjusted dynamically according to the network size and user demand. Secondly, based on the community characteristics, the concept of fuzzy subordinate degree is introduced, then three kinds of community structure mining algorithms are designed: the fuzzy subordinate degree-based algorithm, the improved Kernighan-Lin algorithm, and the enhanced label propagation algorithm. At last, according to the level of privacy, different anonymous graph construction algorithms based on community structure are designed. Furthermore, the simulation experiments show that the three methods of community division can divide the network community effectively. They can be utilized at different privacy levels. In addition, the scheme can satisfy the privacy requirement with minor changes.

Abstract:The differential privacy k -means (DP k -means) clustering algorithm emerged to address the privacy protection challenges in the field of data mining. However, the algorithm encounters difficulties in achieving clustering usability and convergence. Privacy budget ( ε ), a critical parameter determining the noise addition in differential privacy algorithms, garners significant attention. Consequently, researchers have shifted their focus to studying privacy budget allocation strategies within the DP k -means clustering algorithm. However, the selection of a privacy budget allocation strategy in the DP k -means algorithm is an NP-hard problem. Our initial intuition is that genetic algorithms can efficiently discover relatively optimal privacy budget sequences. In this context, we propose a genetic algorithm-based privacy budget allocation strategy (GAPBAS) to ensure the convergence and usability of the DP k -means algorithm. Firstly, convergence is ensured by selecting improved initial centroids and rigorously controlling the minimum privacy budget for the DP k -means algorithm. Additionally, the privacy budget allocation strategy of the DP k -means algorithm is reformulated as a combinatorial optimization problem. This entails merging privacy budgets from multiple iterative rounds into a sequential sequence and utilizing a genetic algorithm to select the optimal privacy budget allocation strategy, thereby significantly enhancing the usability of the DP k -means algorithm. Comparative experiments against the other four privacy budget allocation strategies in the DP k -means algorithm demonstrate the superior performance of the genetic algorithm-based privacy budget allocation strategy at the same level of privacy protection.

Abstract:The privacy-preserving data publishing (PPDP) problem has gained substantial attention from research communities, industries, and governments due to the increasing requirements for data publishing and concerns about data privacy. However, achieving a balance between preserving privacy and maintaining data quality remains a challenging task in PPDP. This paper presents an information-driven distributed genetic algorithm (ID-DGA) that aims to achieve optimal anonymization through attribute generalization and record suppression. The proposed algorithm incorporates various components, including an information-driven crossover operator, an information-driven mutation operator, an information-driven improvement operator, and a two-dimensional selection operator. Furthermore, a distributed population model is utilized to improve population diversity while reducing the running time. Experimental results confirm the superiority of ID-DGA in terms of solution accuracy, convergence speed, and the effectiveness of all the proposed components.

A Two-Dimensional Genetic Algorithm for Identifying Overlapping Communities in Dynamic Networks

Abstract:The analysis of communities and their evolution in dynamic networks is a challenging research with broad applications. The recent studies have found that the overlaps between communities are more densely connected than the non-overlapping parts in some real networks. The findings are different from the present concepts of the overlapping communities. Existing methods may fail to detect this kind of communities. In this paper, we first extend the findings to analyze dynamic networks and develop an effective algorithm for detecting dense overlapping communities and their evolution in a unified process by using evolutionary clustering. We also introduce genetic algorithm with multidimensional chromosome to describe nodes belonging to multiple communities in our framework. The experimental studies demonstrate that our method successfully captures dense overlaps and identifies relevant communities more accurately than the state-of-the-art methods in dynamic networks.

Abstract:Community structure identification has been an important research topic in complex networks and there has been many algorithms proposed so far to detect community structures in complex networks, where most of the algorithms are not suitable for very large networks because of their time-complexity. Genetic algorithm for detecting communities in complex networks, which is based on optimizing network modularity using genetic algorithm, is presented here. It is scalable to very large networks and does not need any priori knowledge about number of communities or any threshold value. It has O(e) time-complexity where e is the number of edges in the network. Its accuracy is tested with the known Zachary Karate Club and College Football datasets. Enron e-mail dataset is used for scalability test.

Abstract:Location privacy preserving is attracting more and more attentions with the wide use of accurate positioning devices. Two kinds of methods based on k-anonymity have been proposed for location privacy preserving. One is spatial cloaking and the other is dummy generation. However, simple cloaking may result in large cloaking region, especially when user distribution is sparse. Large cloaking region means low efficiency and high time cost. Dummy generation will also arouse great extra system cost. In this paper, we propose an approach that combines the two techniques to achieve an ideal complement. On one hand, cloaking algorithm is used to blur precise location into a region so that location privacy can be well protected. On the other hand, to those users whose cloaking region is large, generating limited number of dummies can help decrease the size of region. The effectiveness of our methods has been demonstrated by comprehensive experiments. © Springer-Verlag 2012.

Abstract:There is a surge of community detection on complex network analysis in recent years, since communities often play special roles in the network systems. However, many community structures are overlapping in real word. For example, a professor collaborates with researchers in different fields. In this paper, we propose a novel algorithm to discover overlapping communities. Different from conventional algorithms based on node clustering, our algorithm is based on edge clustering. Since edges usually represent unique relations among nodes, edge clustering will discover groups of edges that have the same characteristics. Thus nodes naturally belong to multiple communities. The proposed algorithm apply a novel genetic algorithm to cluster on edges. A scalable encoding schema is designed and the number of communities can be automatically determined. Experiments on both artificial networks and real networks validate the effectiveness and efficiency of the algorithm.
