Abstract:Fault-tolerant real-time scheduling algorithm is one of the most important means to ensure the timeliness and high availability characteristics of fault-tolerant real-time systems. Existing scheduling models for periodic real-time task in heterogeneous platforms typically require the number of processors in the systems to be determined in advance; hence prohibit the scalability and the performance of distributed systems. The algorithms based on these models also require a large number of schedubility tests which lead to long execution time. To address these problems, we propose a primary and backup replica partition based fault-tolerant scheduling algorithm (PBPFT) based on a scalable scheduling model using heterogeneity that does not have to determine the scale of the distributed system in advance. The PBPFT approach also takes advantage of backup copy overlapping and phasing delay techniques to minimize system redundancy, and adopts the processor grouping technique to simplify algorithm complexity. Comprehensive experiments are conducted, and the results validate high resource utilization and commendable performance of our proposed approach.

Abstract:Big data, cloud computing, and artificial intelligence technologies supported by heterogeneous systems are constantly changing our life and cognition of the world. At the same time, its energy consumption affects the operation cost and system reliability, and this attracts the attention of architecture designers and researchers. In order to solve the problem of energy in heterogeneous system environment, inspired by the results of 0-1 programming, a scheduling method of heuristic and greedy energy saving (HGES) approach is proposed to allocate tasks reasonably to achieve the purpose of energy saving. Firstly, all tasks are assigned to each GPU in the system, and then the tasks are divided into high-value tasks and low-value tasks by the calculated average time value and variance value of all tasks. By using the greedy method, the high-value tasks are assigned first, and then the low-value tasks are allocated. In order to verify the effectiveness and rationality of HGES, different tasks with different inputs and different comparison methods are designed and tested. The experimental results on different platforms show that the HGES has better energy saving than that of existing method and can get result faster than that of the 0-1 programming.

Communication-Efficient Task Scheduling for Real-Time Distributed Computing.

Abstract:In the distributed big data real-time computing platform, the task scheduling has significant impact on the real-time performance. In this paper, we first reveal the inefficiency of the conventional real-time streaming processing scheduling algorithm in the well-known Storm framework. Based on our observations, we propose a communication-efficient task scheduling algorithm taking both physical cluster's computation and communication capacities into consideration. Our goal is to minimize the communication cost under taking full advantage of cluster computing capacity. Due to the non-convex constraints in our problem, we relax the binary integer to a continuous interval so that the condition can meet to handle the $l_{0}$-norm constraint. By introducing an auxiliary variable and constructing penalty function, $l_{0}$-norm can be transformed to obtain a solution for the relaxed problem. In view of the bipartite graph property of our model, we round the fractional solution of the relaxed problem to the integer solution in its sub-graphs to approach the solution of the original problem. Finally, to evaluate the proposed method, we compare it with two conventional scheduling algorithms, which demonstrates that the proposed algorithm outperforms the other two baseline schemes.

Abstract:The multi-task federated learning (FL) problem in the wireless communication system is investigated in this paper. The base station (BS) and wireless users cooperatively perform a two-task FL algorithm in the established model. Users use their local datasets to train two local models of two different tasks. The trained local model of only one task is transmitted to the BS at each time and the BS aggregates the obtained models to calculate a global model, which will be sent back to all users. Since the resources for wireless transmission, such as transmit power and number of subcarriers are limited, the BS have to allocate resources reasonably to minimize the time consumption of the FL procedure while meeting the required learning performance. On the other hand, users are dynamically arranged to participate in different tasks in each iteration. This resource allocation and users arrangement problem is formulated as an optimization problem which aims to minimize time consumption of the two-task FL procedure. To address this nonconvex problem, we first decompose it into two convex sub-problems. Then we propose an iterative algorithm to solve this problem via iteratively obtaining the optimal solution of the joint power control and communication round optimization subproblem, and user arrangement subproblem. Simulation results of this multi-task FL system show that the proposed algorithm can reduce 7.02% and 9.67% completion time compared to the uniform and random user selection schemes respectively.

Abstract:The distributed energy power system needs to provide sufficient and flexible computing power on demand to meet the increasing digitization and intelligence requirements of the smart grid. However, the current distribution of the computing power and loads in the energy system is unbalanced, with data center loads continuously increasing, while there is a large amount of idle computing power at the edge. Meanwhile, there are a large number of real-time computing tasks in the distributed energy power system, which have strict requirements on execution deadlines and require reasonable scheduling of multi-level heterogeneous computing power to meet real-time computing demands. Based on the aforementioned background and issues, this paper studies the real-time service scheduling problem in a multi-level heterogeneous computing network of distributed energy power systems. Specifically, we consider the divisibility of tasks in the model. This paper presents a hierarchical real-time task-scheduling framework specifically designed for distributed energy power systems. The framework utilizes an orchestrating agent (OA) as the execution environment for the scheduling module. Building on this, we propose a hierarchical selection algorithm for choosing the appropriate network layer for real-time tasks. Further, we develop two scheduling algorithms based on greedy strategy and genetic algorithm, respectively, to effectively schedule tasks. Experiments show that the proposed algorithms have a superior success rate in scheduling compared to other current algorithms.

Abstract:Edge computing is a popular paradigm in solving the problems of long time delay and high energy consumption in Internet of Things (IoT) network, which can effectively realize the IoT task offloading by collaboration of multiple edge servers. Nevertheless, how to choose the appropriate edge servers for offloading the dependent subtasks is still a big challenge, considering the limited resources and computing power of the edge servers as well as the start and end execution time of each subtask. These factors have a great impact on the execution efficiency of the whole task. At present, most of the research works focus on single-hop or multi-hop task offloading, where the edge servers farther away are not considered in the offloading decision. Such task offloading strategy is not optimal, and difficult to achieve high parallel execution of tasks, resulting in some delay-sensitive tasks not being completed within the specified time. In this article, a two-stage optimization method is proposed to solve the resource allocation problem between edge servers and tasks. In the first stage, we group tasks according to their priorities, and the group with a higher priority is given the preference to resource allocation, thereby ensuring the timeliness of delay-sensitive tasks. Within the same group, resources are competed according to the game theory, and the total delay of all tasks is optimized. In the second stage, we aim to optimize the energy consumption of each task without increasing its completion time by allocating the computing resources to its subtasks based on their maximum completion time. For group resource allocation, we propose a spatial index tree to store the information of all edge servers for optimal server selection. During the selection process, an online learning based double prediction model is utilized to reduce the energy consumption caused by information transmission. We have evaluated the performance of the experiment on iFogSim simulator, and the experimental results show that our proposed method can achieve better performance in terms of time delay and energy consumption.

Energy-Aware Task Allocation for Large Task Sets on Heterogeneous Multiprocessor Systems

Abstract:In recent decades, the research of energy-aware scheduling on heterogeneous multiprocessor systems is becoming more and more popular. A classic method for real-time task allocation is Linear Programming (LP). However, existing LP formulations are usually regarded as ineffective in solving large-scale allocation problems due to the unacceptable time consumption. In this work, we propose two integer linear programming (ILP) formulations to deal with the allocation problems for large task sets. One exact ILP(1) is formulated to derive an intermediate solution, and the other relaxed ILP(2) is considered to calculate the desired minimum energy. Then the desired minimum energy can be taken as a reference to evaluate the optimality of the intermediate solution. Experimental results on randomly generated task sets demonstrate that our method achieves average 19.2% less energy within limited time than the classic greedy and the state-of-the-art heuristic algorithm.

Abstract:The ubiquity of mobile devices creates a rapidly growing market for mobile applications. Many of these applications involve complex processing tasks that are difficult to run on resource constrained mobile devices. This leads to the emergence of mobile cloud computing, in which cloud-based resources are used to enhance the computing capabilities of mobile devices. In this paper, we consider heterogeneous wireless networks in which multiple resource-rich computing nodes can be used as mobile clouds, and mobile devices can upload computation extensive tasks to these mobile clouds. The goal is to minimize the average task response time through determining whether to upload a task, and to which cloud the task should be uploaded. We formalize this task allocation problem, which is proved to be a NP-hard problem, and propose both offline centralized approach and online distributed approach to address this problem. Simulation results show that our approaches outperform others in terms of task response time in various scenarios.

Abstract:Computation-intensive mobile applications are explosively increasing and cause computation overload for smart mobile devices (SMDs). With the assistance of mobile edge computing and mobile cloud computing, SMDs can rent computation resources and offload the computation-intensive applications to edge clouds and remote clouds, which reduces the application completion delay and energy consumption of SMDs. In this paper, we consider the mobile applications with task call graphs and investigate the task offloading and resource scheduling problem in hybrid edge-cloud networks. Due to the interdependency of tasks, time-varying wireless channels, and stochastic available computation resources in the hybrid edge-cloud networks, it is challenging to make task offloading decisions and schedule computation frequencies to minimize the weighted sum of energy, time, and rent cost (ETRC). To address this issue, we propose two efficient algorithms under different conditions of system information. Specifically, with full system information, the task offloading and resource scheduling decisions are determined based on semidefinite relaxation and dual decomposition methods. With partial system information, we propose a deep reinforcement learning framework, where the future system information is inferred by long short-term memory networks. The discrete offloading decisions and continuous computation frequencies are learned by a modified deep deterministic policy gradient algorithm. Extensive simulations evaluate the convergence performance of ETRC with various system parameters. Simulation results also validate the superiority of the proposed task offloading and resource scheduling algorithms over baseline schemes.
A Task Level-Aware Scheduling Algorithm for Energy Consumption Constrained Parallel Applications on Heterogeneous Computing Systems

Abstract:Energy consumption is a significant concern for both small-scale embedded devices to large-scale data centers. The problem of minimizing the scheduling length of parallel applications with energy constraints in heterogeneous computing systems has garnered widespread attention. The crux of this problem lies in the rational conversion of energy constraints of the application to the energy constraints of each task, utilizing dynamic voltage and frequency scaling (DVFS) technology. To determine the energy constraints of each task, the commonly used method is the task energy pre-allocation strategy. Previous studies only focused on energy allocation for individual tasks, neglecting the consideration of task levels. However, an equitable energy allocation for each task is not necessarily the optimal approach. If the levels of tasks in energy allocation are taken into account, more energy can be allocated to tasks that have a greater impact on the overall application scheduling time, thus effectively reducing the application scheduling time. Therefore, we have proposed a task level-aware scheduling algorithm that allocates energy to each level based on the proportion of the minimum energy consumption for the level, then, the algorithm assigns energy to each task based on the proportion of the task's weighted time in the current level. Extensive experimental results demonstrate that our approach allocates energy reasonably and achieves better performance, effectively reducing the application's schedule length.

Abstract:Cloud computing has become an important paradigm in which scalable resources such as CPU, memory, disk and IO devices can be provided to users to remotely process their applications. In a cloud computing platform, energy consumption accounts for a significant cost portion. This article thus aims to present an energy-efficient scheduling algorithm for processing a user application with a real-time requirement. This problem is formulated as a non-linear mixed integer programming problem. We start with providing an optimal closed-form solution to its relaxation problem that aims to minimize the energy consumption without considering real-time requirements. To meet real-time requirements, we propose how to adjust task placement and resource allocation by making a good tradeoff between energy consumption and task execution time. Lastly, we find two equivalent optimal resource allocation strategies once task placement has been done. We then propose to adjust the start time of task execution such that an application's completion time can be further shortened. Experimental results on two real-case enchmarks and extensive synthetic applications demonstrate that our proposed method finds a schedule that generally has 30 and 20 percent less energy consumption than enhancement heterogeneous earliest finish time (E-HEFT) and genetic algorithm, respectively. Besides, the proposed method has a higher rate to successfully find a feasible schedule than them, and its computation time is close to E-HEFT's, but far less than the genetic algorithm's.

Abstract:In heterogeneous reconfigurable systems including FPGA and CPU, besides software tasks and hardware tasks, there exist hybrid tasks which can be either executed on CPU as software tasks or implemented on FPGA as hardware tasks. This paper mainly focuses on the online scheduling problem within heterogeneous reconfigurable systems. According to a reconfigurable system prototype, a task scheduler model and its corresponding scheduling algorithm are presented. The model combines task allocation and task placement with task migration, making use of the great flexibility of hybrid tasks. Simulation results have demonstrated that the proposed algorithm can provide preferable scheduling performance and reduce the rejection rate.

Abstract:SummaryThe continually increasing energy consumption represents a critical issue in modern heterogeneous computing systems. With the aid of dynamic voltage frequency scaling (DVFS), task scheduling is considered an effective software‐based technique for reducing the total energy consumption and minimizing the overall schedule length (makespan). A natural solution is to reclaim the slack time in a given time‐efficient schedule, which is also referred to as a “two‐pass” method or a “rescheduling” method. A number of studies have focused on slack reclamation to achieve energy reductions through heuristics; although, these methods offer suboptimal solutions. In this article, the rescheduling optimization problem is formulated as a linear program for minimizing an energy objective function subject to precedence and deadline constraints implied in the given schedule. Two types of decision variables, ie, frequency duty factors and task intervals, are defined to set up the linear model. Consequently, an optimal solution to the problem can be provided in a straightforward manner by a linear programming solver, which suggests that such a rescheduling problem belongs to the P (polynomial time) class. The experimental results show the effectiveness of the proposed approach and demonstrate that the performance is superior to that of other competitive algorithms in terms of both energy saving and runtime efficiency.

Abstract:<p>This paper investigates a mobile edge computing environment for video analysis tasks where edge nodes provide their computation capacities to process the computation intensive tasks submitted by end users. First, we introduce a Cloudlet Assisted Cooperative Task Assignment (CACTA) system that organizes edge nodes that are geographically close to an end user into a cluster to collaboratively work on the user's tasks. It is challenging for the system to find an optimal strategy that assigns workload to edge nodes to meet the user's optimization goal. To address the challenge, this paper proposes multiple algorithms for different situations. Firstly, considering the situation that historical data cannot be obtained, a multi-round allocation algorithm based on EMA prediction is proposed, and the experimental results prove the efficiency and necessity of multiple rounds of transmission. To address the second case of obtaining historical data, this paper introduces a prediction-based dynamic task assignment algorithm that assigns workload to edge nodes in each time slot based on the prediction of their capacities/costs and an empirical optimal allocation strategy which is learned from an offline optimal solution from historical data. Experimental results demonstrate that our proposed algorithm achieves significantly higher performance than several other algorithms, and especially its performance is very close to that of an offline optimal solution. Finally, we propose an online task assignment algorithm based on Q-learning, which uses the model-free Q-learning algorithm to actively learn the allocation strategy of the system, and the experimental results verify the superiority and effectiveness of this algorithm.</p>

Abstract:Edge computing has changed the landscape of telecommunication networks. Different from cloud computing in which thousands of servers are centralized in a remote site, computation and storage resources are deployed at the network edge in edge computing, reducing the end-to-end latency and the amount of transmitting data in metro/backbone networks significantly. Due to the limited resource capacity in a single edge node and the requirements of distributed applications, some applications are supposed to be decomposed into multiple interdependent tasks and executed in distributed resource-constrained nodes. Assigning tasks to geographically distributed edge nodes is quite challenging because of the allocation of multidimensional resources (i.e., computation, storage, and transmission) as well as constraints of the interdependency between different tasks. Strategies that take only one factor into account for optimization will cause improper task assignments, leading to higher end-to-end latency and lower resource utilization efficiency. To solve this problem, we formulate a mathematical model aiming at minimizing the job completion time by jointly considering the availability of multidimensional resources and the interdependency among different tasks. We obtain optimal results in small topology by using optimization software that validates the correctness of the proposed mathematical model. Furthermore, we analyze the complexity and design of a practical algorithm by narrowing the searching space in large-scale topology. Simulation results present its effectiveness over greedy algorithms. Finally, we conduct a proof-of-concept experiment to validate the feasibility of the proposed strategy.

Abstract:Along with the growth of computing requirements, edge devices, such as satellites and unmanned aerial vehicles, are equipped with heterogeneous multiprocessor systems to cope with complicated missions, including attitude control, signal processing, and objective detection. Concerning the extremely limited power on these devices, reducing the energy and time overhead of task execution evolves into a crucial challenge. Therefore, a multiobjective energy-efficient task scheduling technique (METSM) is proposed. First, a mathematical model is established for the energy-efficient task scheduling problem on edge heterogeneous multiprocessor systems. In this model, both makespan and total energy consumption are the optimization objectives. The decision variables include the task execution sequence, processor assignment, and dynamic voltage and frequency scaling level for each processor. Second, a problem-specific algorithm, namely, iterated greedy-based multiobjective optimizer (IMO), is proposed. Specifically, destruction-reconstruction and local search are redesigned for optimizing task scheduling and resource allocation. Considering local optima avoidance, a probabilistic mutation operation is developed. In addition, multiobjective-oriented strategies of optimal solution selection and acceptance criteria are adopted to accelerate the convergence. Finally, our proposed IMO is compared with several of the latest algorithms through multiple performance metrics. The experimental results show that IMO can obtain optimal Pareto fronts among several multiobjective methods. Savings of approximately 10% and 12% in time and power consumption, respectively, can be achieved by IMO. Moreover, in comparison with classic list-based heuristics for solving test cases, while IMO maintains a similar makespan, energy is reduced by nearly 90%.

Abstract:With the development of computationally intensive applications, the demand for edge cloud computing systems has increased, creating significant challenges for edge cloud computing networks. In this paper, we consider a simple three-tier computational model for multiuser mobile edge computing (MEC) and introduce two major problems of task scheduling for federated learning in MEC environments: (1) the transmission power allocation (PA) problem, and (2) the dual decision-making problems of joint request offloading and computational resource scheduling (JRORS). At the same time, we factor in server pricing and task completion, in order to improve the user-friendliness and fairness in scheduling decisions. The solving of these problems simultaneously ensures both scheduling efficiency and system quality of service (QoS), to achieve a balance between efficiency and user satisfaction. Then, we propose an adaptive greedy dingo optimization algorithm (AGDOA) based on greedy policies and parameter adaptation to solve the PA problem and construct a binary salp swarm algorithm (BSSA) that introduces binary coding to solve the discrete JRORS problem. Finally, simulations were conducted to verify the better performance compared to the traditional algorithms. The proposed algorithm improved the convergence speed of the algorithm in terms of scheduling efficiency, improved the system response rate, and found solutions with a lower energy consumption. In addition, the search results had a higher fairness and system welfare in terms of system quality of service.
Energy-Efficient Real-Time Task Allocation in a Data Center.

Abstract:Energy saving is one of the most important issues in the design of data centers. Dynamic Voltage and Frequency Scaling (DVFS) is recognized as an effective technique for achieving the tradeoff between system performance and energy saving. Many previous works addressed the DVFS-based energy-aware task allocation using total workload (execution time) of tasks, but it is extremely difficult to obtain in some scenarios. In this paper, we investigate the task allocation to minimize the energy consumption of clusters based on a new common task model, which present task requirements using the minimum frequency instead of execution time. We propose Energy Consumption Ratio (ECR) to evaluate the energy consumption of executing a task under different frequencies, which are constants to processors. Thus, the energy efficient task allocation problem can be converted into minimizing the total ECR. We proved this optimization problem is analogous but more difficult than Variable Size Bin Packing. We propose two lower-order polynomial-time heuristics, allocating tasks among servers. Plenty of experiments show that our algorithms outperform some other energy-aware strategies on energy saving. And we also proved our task allocation mechanism do achieve significant energy saving in a real testbed.

Abstract:The scheduling of a many-task workflow in a distributed computing platform is a well known NP-hard problem. The problem is even more complex and challenging when the virtualized clusters are used to execute a large number of tasks in a cloud computing platform. The difficulty lies in satisfying multiple objectives that may be of conflicting nature. For instance, it is difficult to minimize the makespan of many tasks, while reducing the resource cost and preserving the fault tolerance and/or the quality of service (QoS) at the same time. These conflicting requirements and goals are difficult to optimize due to the unknown runtime conditions, such as the availability of the resources and random workload distributions. Instead of taking a very long time to generate an optimal schedule, we propose a new method to generate suboptimal or sufficiently good schedules for smooth multitask workflows on cloud platforms.

Abstract:Cloud–edge heterogeneous network is an emerging technique built on edge infrastructure, which is based on the core of cloud computing technology and edge computing capabilities. The joint problem of computation offloading, cache decision, and resource allocation for cloud–edge heterogeneous network system is a challenging issue. In this article, we investigate the joint problem of computation offloading, cache decision, transmission power allocation, and CPU frequency allocation for cloud–edge heterogeneous network system with multiple independent tasks. The goal is to minimize the weighted sum cost of the execution delay and energy consumption while guaranteeing the transmission power and CPU frequency constraint of the tasks. The constraint of computing resource and cache capacity of each access point (AP) are considered as well. The formulated problem is a mixed-integer nonlinear optimization problem. In order to solve the formulated problem, we propose a two-level alternation method framework based on reinforcement learning (RL) and sequential quadratic programming (SQP). In the upper level, given the allocated transmission power and CPU frequency, the task offloading decision and cache decision problem is solved using the deep -network method. In the lower level, the optimal transmission power and CPU frequency allocation with the offloading decision and cache decision is obtained by using the SQP technique. Simulation results demonstrate that the proposed scheme achieves significant reduction on the sum cost compared to other baselines.
