Self-supervised Learning Advance Fault Diagnosis of Rotating Machinery

Abstract:Although the approach of using a large number of unlabeled data in self-supervised pre-training and followed by a supervised fine-tuning has achieved success in image recognition, it has received limited attention in fault diagnosis and analysis. On one hand, due to the weakness of early features and various unseen failure modes, it is quite hard to get the label of collecting data. On the other hand, under the strong noise environment, the representation of time and frequency features of original vibration signals is important to improve the performance of fault diagnosis. To construct more information of positive pairs for self-supervised learning, a self-supervised fault detection approach named WT-MICLe for mechanical systems is presented in this paper based on Wavelet Transform (WT), Multi-Instance Contrastive Learning (MICLe), and Residual Neural Network (ResNet). To begin with, WT is applied to extracting features from original signals. Then, visual representations are constructed for self-supervised learning by using MICLe. We present the proposed self-supervised method for fault diagnosis based on contrastive learning. The experiment is implemented to assess the effectiveness of the approach. With a few labeled data, the results overall have shown that the proposed self-supervised approach for fault diagnosis is robust.
