Abstract:It is a critical issue to reduce the enormous amount of data in the processing, storage and transmission of a hologram in digital format. In photograph compression, the JPEG standard is commonly supported by almost every system and device. It will be favorable if JPEG standard is applicable to hologram compression, with advantages of universal compatibility. However, the reconstructed image from a JPEG compressed hologram suffers from severe quality degradation since some high frequency features in the hologram will be lost during the compression process. In this work, we employ a deep convolutional neural network to reduce the artifacts in a JPEG compressed hologram. Simulation and experimental results reveal that our proposed "JPEG + deep learning" hologram compression scheme can achieve satisfactory reconstruction results for a computer-generated phase-only hologram after compression.

End-to-end Compression-Aware Computer-Generated Holography.

Abstract:Joint photographic experts group (JPEG) compression standard is widely adopted for digital images. However, as JPEG encoding is not designed for holograms, applying it typically leads to severe distortions in holographic projections. In this work, we overcome this problem by taking into account the influence of JPEG compression on hologram generation in an end-to-end fashion. To this end, we introduce a novel approach to merge the process of hologram generation and JPEG compression with one differentiable model, enabling joint optimization via efficient first-order solvers. Our JPEG-aware end-to-end optimized holograms show significant improvements compared to conventional holograms compressed using JPEG standard both in simulation and on experimental display prototype. Specifically, the proposed algorithm shows improvements of 4 dB in peak signal-to-noise ratio (PSNR) and 0.27 in structural similarity (SSIM) metrics, under the same compression rate. When maintained with the same reconstruction quality, our method reduces the size of compressed holograms by about 35% compared to conventional JPEG-compressed holograms. Consistent with simulations, the experimental results further demonstrate that our method is robust to JPEG compression loss. Moreover, our method generates holograms compatible with the JPEG standard, making it friendly to a wide range of commercial software and edge devices.

Abstract:The traditional two-dimensional JND (Just Noticeable Difference) model can only estimate the minimum noticeable difference of the planar image, and is not completely suitable for the large field of view image under virtual stereo vision. First, according to the visual characteristics of the human eye, corresponding binocular observation experiments are designed for the four masking characteristics of brightness, contrast, fovea and stereo depth, and the mathematical model of JND is established through experimental data, and compared with other current JND models. The results show that this model can remove more visual redundancy under the same perceptual quality. Then the visual perception redundancy model is applied to image compression. For this purpose, a multi-level compression algorithm is proposed. The algorithm performs different levels of color level quantization on different regions of the image according to the human eye color difference threshold. The quantization process which combines the Floyd-Steinberg error dithering algorithm can remove visual redundant data. Finally, the algorithm verification is completed on the FPGA (Field-Programmable Gate Array) hardware platform. The results show that the average bit compression rate of the algorithm can reach 61.65 A, which can effectively reduce the amount of transmission data required for VR (Virtual Reality) images.

Abstract:Although it is traditionally believed that lossy image compression, such as JPEG compression, has a negative impact on the performance of deep neural networks (DNNs), it is shown by recent works that well-crafted JPEG compression can actually improve the performance of deep learning (DL). Inspired by this, we propose JPEG-DL, a novel DL framework that prepends any underlying DNN architecture with a trainable JPEG compression layer. To make the quantization operation in JPEG compression trainable, a new differentiable soft quantizer is employed at the JPEG layer, and then the quantization operation and underlying DNN are jointly trained. Extensive experiments show that in comparison with the standard DL, JPEG-DL delivers significant accuracy improvements across various datasets and model architectures while enhancing robustness against adversarial attacks. Particularly, on some fine-grained image classification datasets, JPEG-DL can increase prediction accuracy by as much as 20.9%. DeepN-JPEG: A Deep Neural Network Favorable JPEG-based Image Compression Framework

Abstract:As one of most fascinating machine learning techniques, deep neural network (DNN) has demonstrated excellent performance in various intelligent tasks such as image classification. DNN achieves such performance, to a large extent, by performing expensive training over huge volumes of training data. To reduce the data storage and transfer overhead in smart resource-limited Internet-of-Thing (IoT) systems, effective data compression is a "must-have" feature before transferring real-time produced dataset for training or classification. While there have been many well-known image compression approaches (such as JPEG), we for the first time find that a human-visual based image compression approach such as JPEG compression is not an optimized solution for DNN systems, especially with high compression ratios. To this end, we develop an image compression framework tailored for DNN applications, named "DeepN-JPEG", to embrace the nature of deep cascaded information process mechanism of DNN architecture. Extensive experiments, based on "ImageNet" dataset with various state-of-the-art DNNs, show that "DeepN-JPEG" can achieve ~3.5x higher compression rate over the popular JPEG solution while maintaining the same accuracy level for image recognition, demonstrating its great potential of storage and power efficiency in DNN-based smart IoT system design.

Phase-difference-based Compression of Phase-Only Holograms for Holographic Three-Dimensional Display.

Abstract:In holographic three-dimensional (3D) display, holograms for reconstructing 3D scenes require huge storage space and high transmission bandwidth. Holographic data must be compressed for practical applications. The holograms for 3D display are commonly represented in pure-phase format. Existing hologram compression techniques are generally not designed to handle phase-only holograms. In this paper, we propose a phase-difference-based compression method to compress phase-only holograms for holographic 3D display. Phase-only holograms are decomposed into grayscale images representing the phase distance and binary images containing the sign information of the phase difference. The grayscale images can be better handled by common image compression algorithms since their pixel values are proportional to the phase distance reflecting the distance between complex amplitudes. The binary images are compressed by lossless bi-level image coding. The compressed grayscale images and binary images can be synthesized to recover the phase-only holograms and reconstruct the 3D scenes. The advantages of the proposed method over existing image coding standards are verified by numerical simulations.

Abstract:This paper provides a method to build a deep learning image coding system based on inverse problem, choosing a suitable measurement operator to reduce the amount of information transmitted at the sender, and reconstructing the original image by tackling the inverse problem at the receiver. Unlike most compressed sensing (CS) methods, the proposed coding scheme does not rely on sparsity but uses the structural priors of the generative adversarial networks (GAN) to solve the inverse problem. The proposed model trains the GAN to learn a mapping from the latent space to the sample space formed by correlated images on the cloud. Then the measurements are used to localize the optimal latent variable in the representation space which corresponding to the original image in the sample space. The proposed method encodes and transmits the measurements instead of the original image, which greatly reduces the cost of transmission while ensuring the quality of the reconstructed the image at high compression ratios. To the best of our knowledge, this is the first time to introduce the GAN-based inverse problem in the field of the deep image coding area. The experimental results show that the visual quality of the images generated by the proposed scheme is better than the traditional encoding scheme JPEG2000. Especially in the case of extremely high compression ratios, the proposed scheme can still maintain good performance.

Efficient Learned Lossless JPEG Recompression

Abstract:JPEG is one of the most popular image compression methods. It is beneficial to compress those existing JPEG files without introducing additional distortion. In this paper, we propose a deep learning based method to further compress JPEG images losslessly. Specifically, we propose a Multi-Level Parallel Conditional Modeling (ML-PCM) architecture, which enables parallel decoding in different granularities. First, luma and chroma are processed independently to allow parallel coding. Second, we propose pipeline parallel context model (PPCM) and compressed checkerboard context model (CCCM) for the effective conditional modeling and efficient decoding within luma and chroma components. Our method has much lower latency while achieves better compression ratio compared with previous SOTA. After proper software optimization, we can obtain a good throughput of 57 FPS for 1080P images on NVIDIA T4 GPU. Furthermore, combined with quantization, our approach can also act as a lossy JPEG codec which has obvious advantage over SOTA lossy compression methods in high bit rate (bpp$>0.9$).

Abstract:We proposed a phase retrieval combined with the deep learning denoising method in holographic data storage. By learning the relationship between the captured intensity images and the simulation truth images, the deep learning convolutional neural network can have a good grasp of the complex noise patterns in the captured images. Therefore, we can denoise the single-shot captured image to improve image quality significantly. We used the denoised image to retrieve phase by combining single-shot iterative Fourier transform algorithm. The experiment results showed that the bit error rate can be reduced by 6.7 times using the denoised image, which proved the feasibility of the neural network denoising method in the phase-modulated holographic data storage system. We also analyzed the tolerances of our method to show its practicability.

Abstract:This paper proposes an optical image compression and encryption transmission based on deep learning and ghost imaging, which uses ghost imaging as a point-to-face transmission mode to reduce the influence of chaotic medium and turbulence on the communication channel, and combine with the deep learning to improve the reconstructed image resolution. In this method, first, the image is preprocessed by JPEG to obtain a compressed image, and the compressed image is transmitted as an image to be transmitted, which can improve the transmission rate; then, the ghost imaging is used for transmission, which can improve the anti-interference ability and transmission security of the transmission; finally, the problem of poor image quality after ghost-imaging transmission, using deep learning for reconstruction, which can improve the resolution of the image. In the simulation experiment, feasibility analysis, safety analysis, and robustness analysis were carried out, respectively, and the experimental results were objectively evaluated using correlation methods such as peak signal-to-noise ratio, mutual information, and histogram. The experimental results show that the proposed method can provide a feasible and secure optical communication image transmission method and realize high-resolution transmission image reconstruction, which has guiding significance for optical communication.

Optimized Decoupled Structure with Non-Local Attention for Deep Image Compression

Abstract:Recently, a decoupled framework for learning-based image compression has been proposed and adopted into the JPEG AI image coding standard developed by ISO/IEC WG1. The decoupled structure disentangles the sample reconstruction process and the entropy decoding process, making the decoding extremely fast. The corresponding techniques constitute the essential parts of the JPEG AI verification model software. However, its analysis transform and synthesis transform are relatively simple, which are built with stacked convolution layers, thereby may lack the capability to interpret data correlations. In this work, we enhance the transform networks by introducing the non-local attention mechanism, which has proven efficient in image compression tasks. The proposed framework thus shares the merits of the fast decoding from the decoupled architecture and the strong transform capabilities from the non-local attention, making it a stronger candidate for practical end-to-end image codec deployment. Experimental results on the Kodak test set and JPEG AI CfP test set show that our method achieves better BDRate performance compared to the original Decoupled-anchor and significantly faster decoding speed compared to NIC. The proposed solution has been adopted by the IEEE 1857.11 Working Subgroup (1857.11 WSG) in developing neural network-based image coding standards in the 10th Meeting.
Computer-generated Hologram Compression with Attention-Based Deep Convolutional Neural Network

Abstract:We propose an attention-based deep convolutional neural network for computer generated hologram (CGH) compression, where a channel attention mechanism is applied to both computer generated hologram compression and reconstruction. By applying deep convolutional neural networks in the compression process, we can extract more compact and representative information than bicubic interpolation. Additionally, a channel attention mechanism is applied to selectively emphasize informative features and suppress less useful ones for both CGH compression and reconstruction. By employing attention mechanisms to enhance the feature representation ability of deep convolutional neural networks, we can further improve the performance of the reconstructed computer generated hologram. Experimental results show our method can better recover the compressed computer generated hologram than only employing convolutional neural networks in the reconstruction process.

Abstract:Recent deep learning approaches have shown remarkable promise to enable high fidelity holographic displays. However, lightweight wearable display devices cannot afford the computation demand and energy consumption for hologram generation due to the limited onboard compute capability and battery life. On the other hand, if the computation is conducted entirely remotely on a cloud server, transmitting lossless hologram data is not only challenging but also result in prohibitively high latency and storage. In this work, by distributing the computation and optimizing the transmission, we propose the first framework that jointly generates and compresses high-quality phase-only holograms. Specifically, our framework asymmetrically separates the hologram generation process into high-compute remote encoding (on the server), and low-compute decoding (on the edge) stages. Our encoding enables light weight latent space data, thus faster and efficient transmission to the edge device. With our framework, we observed a reduction of 76% computation and consequently 83% in energy cost on edge devices, compared to the existing hologram generation methods. Our framework is robust to transmission and decoding errors, and approach high image fidelity for as low as 2 bits-per-pixel, and further reduced average bit-rates and decoding time for holographic videos.
Deep Image Compression via End-to-End Learning

Abstract:We present a lossy image compression method based on deep convolutional neural networks (CNNs), which outperforms the existing BPG, WebP, JPEG2000 and JPEG as measured via multi-scale structural similarity (MS-SSIM), at the same bit rate. Currently, most of the CNNs based approaches train the network using a L2 loss between the reconstructions and the ground-truths in the pixel domain, which leads to over-smoothing results and visual quality degradation especially at a very low bit rate. Therefore, we improve the subjective quality with the combination of a perception loss and an adversarial loss additionally. To achieve better rate-distortion optimization (RDO), we also introduce an easy-to-hard transfer learning when adding quantization error and rate constraint. Finally, we evaluate our method on public Kodak and the Test Dataset P/M released by the Computer Vision Lab of ETH Zurich, resulting in averaged 7.81% and 19.1% BD-rate reduction over BPG, respectively.

Abstract:Deep learning presents a highly effective for computer-generated holography (CGH). However, existing learning-based CGH algorithms may encounter significant obstacles in generating high-quality holograms for binary images. This study proposes a novel diffraction model-driven neural network, termed load sharing yielding holography (LSY-Holo), which leverages a dual-branch architecture and a global structural similarity index measure (Global_SSIM) loss function to generate phase-only holograms (POHs). LSY-Holo framework facilitates capturing global information, enhancing the network's performance to address the ill-posed inverse problem. To further optimize the model for binary images, the research introduces a custom Binary dataset alongside a stochastic homogenization preprocessing method (SHPM), which mitigates the prevalent issue of excessive noise in reconstructed images. Additionally, this deep learning approach is integrated with an iterative algorithm, which employs holograms rapidly generated by LSY-Holo as the initial phase of the AdamW Holography (AH) algorithm. This strategy significantly accelerates the convergence of the iterative process. LSY-Holo is further extended to 3D scenes, enabling dynamic defocusing and focusing effects at varying depths. Results from numerical simulations and full-color optical reconstruction experiments demonstrate that the proposed method can enhance image quality and effectively reduce the artifacts in reconstructed images.

Abstract:We present a CodedVision framework to achieve image content understanding and compression jointly, leveraging the recent advances in deep neural networks. We have introduced an eight-layer deep residual network to extract image features for compression and understanding. For compression, a scalar quantizer and an entropy coder are utilized to remove redundancy. Rate-distortion optimization is integrated to improve the coding efficiency where rate is estimated via a piecewise linear approximation. A noticeable 7.8% BD-Rate (Bjontegaard delta rate) gain is presented against the state-of-the-art HEVC intra based image compression. For content understanding, we patch another residual network-based classifier to perform the classification, with reasonable accuracy at the current stage.
Unified learning-based lossy and lossless JPEG recompression

Abstract:JPEG is still the most widely used image compression algorithm. Most image compression algorithms only consider uncompressed original image, while ignoring a large number of already existing JPEG images. Recently, JPEG recompression approaches have been proposed to further reduce the size of JPEG files. However, those methods only consider JPEG lossless recompression, which is just a special case of the rate-distortion theorem. In this paper, we propose a unified lossly and lossless JPEG recompression framework, which consists of learned quantization table and Markovian hierarchical variational autoencoders. Experiments show that our method can achieve arbitrarily low distortion when the bitrate is close to the upper bound, namely the bitrate of the lossless compression model. To the best of our knowledge, this is the first learned method that bridges the gap between lossy and lossless recompression of JPEG images.

The JPEG Pleno Learning-based Point Cloud Coding Standard: Serving Man and Machine

Abstract:Efficient point cloud coding has become increasingly critical for multiple applications such as virtual reality, autonomous driving, and digital twin systems, where rich and interactive 3D data representations may functionally make the difference. Deep learning has emerged as a powerful tool in this domain, offering advanced techniques for compressing point clouds more efficiently than conventional coding methods while also allowing effective computer vision tasks performed in the compressed domain thus, for the first time, making available a common compressed visual representation effective for both man and machine. Taking advantage of this potential, JPEG has recently finalized the JPEG Pleno Learning-based Point Cloud Coding (PCC) standard offering efficient lossy coding of static point clouds, targeting both human visualization and machine processing by leveraging deep learning models for geometry and color coding. The geometry is processed directly in its original 3D form using sparse convolutional neural networks, while the color data is projected onto 2D images and encoded using the also learning-based JPEG AI standard. The goal of this paper is to provide a complete technical description of the JPEG PCC standard, along with a thorough benchmarking of its performance against the state-of-the-art, while highlighting its main strengths and weaknesses. In terms of compression performance, JPEG PCC outperforms the conventional MPEG PCC standards, especially in geometry coding, achieving significant rate reductions. Color compression performance is less competitive but this is overcome by the power of a full learning-based coding framework for both geometry and color and the associated effective compressed domain processing.

Abstract:Learning-based image compression has raised increasing interests in the last few years. Currently, Joint Photographic Experts Group (JPEG) is working on the standardization of learning-based image compression as JPEG AI. It adopts a deep neural network based encoder-decoder architecture with hyperprior based probability formulation for entropy coding. JPEG AI currently contains two coding profiles: Base Operating Point (BaseOP) and High Operating Point (HighOP). Among the various techniques developed in JPEG AI, Multistage Context Model (MCM) was adopted as the context model to perform intra prediction in HighOP. It transforms the spatially progressive context prediction into sub-image feature prediction among channels via feature down-shuffling. However, in this prediction process, sub-image features are not spatially aligned to each other, and directly using the neighboring sub-image features cannot provide accurate prediction. Moreover, the distributions of residual features generated by MCM are also not consistent with that of the hyper scale decoder, which is used to construct the probability model in the entropy coding of residual features, leading to suboptimal residual coding. To address the above problems, we propose an Aligned Intra Prediction (AIP) and Aligned Hyper Scale Decoder (AHSD) under MCM for JPEG AI coding. AIP aligns the reference sub-image features to the to-be-predicted feature in MCM. AHSD further generates hyper scale features with matched distributions to the residual features. Experimental results demonstrate that the proposed method improves the coding performance by 1.3% in terms of BD-rate saving over the JPEG AI reference software.

Ultra High Fidelity Deep Image Decompression With l∞-Constrained Compression

Abstract:We propose a novel asymmetric image compression system of light l∞ -constrained predictive encoding and heavy-duty CNN-based soft decoding. The system achieves superior rate-distortion performances over the best of existing image compression methods, including BPG, WebP, FLIF and recent CNN codecs, in both l2 and l∞ error metrics, for bit rates near or above the threshold of perceptually transparent reconstruction. These remarkable coding gains are made by deep learning for compression artifact removal. A restoration CNN is designed to map a lossy compressed image to its original. Its unique strength is to enforce a tight error bound on a per pixel basis. As such, no small distinctive structures of the original image can be dropped or distorted, even if they are statistical outliers that are otherwise sacrificed by mainstream CNN restoration methods.
