Abstract:With the rapid development of spaceborne synthetic aperture radar (SAR) technology and the acquisition of a large volume of SAR images, SAR image interpretation has become an urgent and difficult research topic. SAR image statistical modeling is one of the theoretical foundations for SAR image interpretation. It is of great value for the in-depth analysis of SAR images. This article reviews the major developments of SAR image statistical modeling since its beginning, including more than 20 statistical distributions of eight statistical models, and gives their derivations and expressions, which can be used as a basic reference for the statistical modeling of SAR images (see "Notations and Definitions").

Abstract:Following on the first part of our review of synthetic aperture radar (SAR) image statistical modeling [1], which concerns single-pixel statistical models, this article extends our discussion to spatial correlation analysis, focusing on SAR spatial correlation models and SAR clutter simulation methods. Two types of spatial correlation models, the product model and the coherent scatterer model, are summarized: the first considers correlation characteristics from the image itself while the second analyzes spatial correlation stemming from the underlying scatterer and the physical imaging process. In addition, we review four spatially correlated clutter simulation methods based on two classical distributions (K and G°): a product model-based method, an inverse transform method (ITM)-based approach, a coherent scatterer model-based technique, and the generalized Gaussian coherent scatterer (GGCS) approach. We discuss the advantages and disadvantages of these models and methods and provide references for further research into the statistical modeling of SAR images.

Abstract:SAR image due to its nature of coherent imaging manifests both deterministic semantic information and speckle-like statistical textures. It is necessary to have a general representation scheme of the semantic-statistical two-layer hierarchy of SAR image so that semantic and textural information can be separated. Inspired by the correlated clutter simulation method proposed by Bustos et al [1-2], this paper studies a semantic-statistical convolution scheme to generate a SAR image from a semantic map. For each terrain type, we estimate the intensity distribution and correlated texture model and then generate textures with correlated clutter. The method is tested on actual SAR images of E-SAR data including urban and forest areas and Flevoland AirSAR data with 15 terrains.

Abstract:Pixel-level remote sensing image time series retain more raw information and detail level information on surface features.It contributes to extract feature information more accurately and reveal the surface change rules.Aimed at SAR image data set,this paper presented the modeling method of pixel-level SAR image time series,the main procedure of which includes radiometric correction and high-precision geometric registration.The method transforms SAR images stacked data into time series textual data consisting of discrete backscattering coefficients.21wide-swath ENVISAT ASAR images from 2006to 2009which have 150mresolution with a pixel spacing of 75mwere utilized to model pixel-level SAR image time series.Geometric accuracy and radiometric accuracy were evaluated respectively in the experiment.The experimental results showed that the modeling method possesses high precision both in geometry and radiation and applied to identify the ground object type.It will play a unique advantage in features extraction,clustering analysis and change detection,bearing strong potential in application.
Comparative Analysis of Statistical Characteristics Between Bi-SAR Images and Mon-SAR Images

Abstract:The transmitter and receiver of bistatic SAR (Synthetic Aperture Radar) are placed on two different carrier platforms, which provide higher flexibility and have become one of the research hotspots in the field of SAR. Compared to monostatic SAR, bistatic SAR has many unique advantages. Due to the misalignment of the bistatic SAR transmitter and receiver, there are differences in imaging results between bistatic SAR and monostatic SAR. SAR image interpretation is key to the application of SAR images, and accurately describing the characteristics of SAR images is a prerequisite for effectively understanding SAR images. In order to observe the differences in statistical characteristics between the two, in this paper, we use statistical modeling methods to compare and analyze the texture characteristics of SAR images. Firstly, some texture SAR images were selected, and then the generalized Gamma distribution model from the empirical model was used to statistically model the bistatic SAR and monostatic SAR images. The parameter decoupling method was used to effectively estimate the model parameters. Finally, the local variation coefficient, which describes scene heterogeneity, was calculated to measure the texture information of the images. By processing the measured data, we found that, for the same imaging scene, monostatic SAR imaging results have stronger texture information compared to bistatic SAR. This article analyzes the differences in image characteristics between bistatic SAR and monostatic SAR from the perspective of statistical characteristics, laying the foundation for SAR image interpretation and target recognition.
SAR to Optical Image Translation with Color Supervised Diffusion Model

Abstract:Synthetic Aperture Radar (SAR) offers all-weather, high-resolution imaging capabilities, but its complex imaging mechanism often poses challenges for interpretation. In response to these limitations, this paper introduces an innovative generative model designed to transform SAR images into more intelligible optical images, thereby enhancing the interpretability of SAR images. Specifically, our model backbone is based on the recent diffusion models, which have powerful generative capabilities. We employ SAR images as conditional guides in the sampling process and integrate color supervision to counteract color shift issues effectively. We conducted experiments on the SEN12 dataset and employed quantitative evaluations using peak signal-to-noise ratio, structural similarity, and fréchet inception distance. The results demonstrate that our model not only surpasses previous methods in quantitative assessments but also significantly enhances the visual quality of the generated images.

Abstract:Superpixel based SAR image classification methods can take advantage of the contextual information in SAR images effectively, leading to robust classification results. The accuracy of superpixel generation has great impact on the performance of the following classification stage. In this paper, based on the property of SAR images, an energy minimizing based superpixel generation approach is proposed for SAR images. The energy function is composed of two parts. The data term is defined according to the statistical characteristic of SAR images, and the regularization term is defined by using the ratio of mean intensity. Then the superpixel generation is performed by energy minimizing with graph cut based energy minimization method. Experimental results on both synthetic and real SAR image data verify the good performance of the proposed approach. Compared with several superpixel approaches, the proposed approach can deal with speckle noise more effectively, resulting in better applicability for SAR images.
A Variational Level Set SAR Image Segmentation Approach Based on Statistical Model

Abstract:SAR image automatic segmentation is a hard work due to the presence of speckle noise. In this paper, a variational level set approach for SAR image is presented. A new energy functional is defined by taking account of a statistical model of speckle noise. The energy functional is with respect to level set function, which is obviously different from the energy functional with respect to parameterized curve in general level set approach. Segmentation is implemented by minimizing the energy formulation via level set approach. The performance of the approach is verified by MSTAR SAR images. It shows that the energy well describes the property of SAR image, thus accurately and automatically extracts the regions of interest in SAR image but without any speckle pre-processing step.
Amplitude and Texture Feature Based Sar Image Classification with A Two-Stage Approach

Abstract:This paper presents an SAR image classification approach that takes advantage of both amplitude and texture features. The proposed approach is based on superpixels obtained with some over-segmentation methods, and consists of two stages. In the first stage, the SAR image is classified with amplitude and texture feature used separately. Specifically, we use statistical model based maximum-likelihood method for amplitude based classification. Meanwhile, we classify the SAR image with the support vector machine (SVM) method by taking histograms generated with sparse coded morphological profiles as feature. To combine classification results produced with amplitude and texture features, a second refine stage is proposed based on the conditional random field (CRF) method. We define the CRF based on region adjacent graph (RAG) of superpixels. The unary term of the CRF is based on fusing classification scores produced by two classifiers in the first stage. Therefore, both of amplitude and texture information are used for the final classification. The graph cut (GC) algorithm is used to optimize the CRF model. We show experimental results on real SAR data, which verify the effectiveness of the proposed approach.

Abstract:Urban area man-made target detection based on SAR images has been a challenging field for years due to the complicated scattering mechanisms of dense buildings and the poor visual quality of SAR images caused by speckle noises. To overcome the effect of speckle noise, a substantial portion of SAR image processing methods are based on statistical characteristics. In this paper, the importance of using non-zero mean models is discussed in the experiments, and two statistical models are proposed for polarization SAR image processing. Moreover, a non-zero mean index is invented to test the scattering determinacy level. This work will be very helpful for the improvement of urban area information extraction based on fully polarized SAR images.

Abstract:In this paper, a new method is proposed for unsupervised speckle level estimation in synthetic aperture radar (SAR) images. It is assumed that fully developed speckle intensity has a Gamma distribution. Based on this assumption, estimation of the equivalent number of looks (ENL) is transformed into noise variance estimation in the logarithmic SAR image domain. In order to improve estimation accuracy, texture analysis is also applied to exclude areas where speckle is not fully developed (e.g., urban areas). Finally, the noise variance is estimated by a 2-dimensional autoregressive (AR) model. Abstract:The development of SAR technology brings a large number of high-resolution SAR images. SAR clutter in these images contains rich environmental information which is inappropriate to be modeled by a single simple statistical model as traditional approaches. It is very critical to reveal the physical information stored in these images for further interpretation and applications of SAR images. This paper aims to give a physical perspective of the correlated SAR clutter starting from the coherent scatterer model. The Gaussian coherent scatterer (GGCS) model kicks off the first step in modeling the physical processes of clutter and the probabilistic graphical network is expected to be an effective intelligent realization of the GGCS model.

Abstract:To overcome the problems of large data volumes and strong speckle noise in synthetic aperture radar (SAR) images, a multi-scale level set approach for SAR image segmentation is proposed in this article. Because the multi-scale analysis of SAR images preserves their highest resolution features while additionally making use of sets of images at lower resolutions to improve specific functions, the proposed method is useful for removing the influence of speckle and, at the same time, preserving important structural information. The Gamma distribution is one of the most commonly used models employed to represent the statistical characteristics of speckle noise in a SAR image and it is introduced to define the energy functional. Moreover, based on the multi-scale level set framework, an improved multi-layer approach is introduced for multi-region segmentation. To obtain a fast and more accurate result, a novel threshold segmentation result is used to represent the initial segmentation curve. The experiments with synthetic and real SAR images demonstrate the effectiveness of the new method.

Abstract:Visual interpretation of SAR images plays a critical role in remote sensing applications. For rapidly obtaining the image suitable for human observation, a new method of visualization for SAR images is proposed in this paper. The statistics of the SAR data, including the single channel data intensity and the span of the Pol-SAR data, are derived. The proposed method is a parameterized method based on the characteristic statistic of the SAR data. Using the AIRSAR data, the effectiveness of the proposed method is demonstrated by comparing to the traditional algorithm.

Abstract:A signal-model-based SAR image formation algorithm is proposed in this paper. A model is used to describe the received signal, and each scatterer can be characterized by a set of its parameters. Two parameter estimation methods via atomic decomposition are presented: ( 1) applying 1-D matching pursuit to azimuthal projection data; ( 2) applying 2-D matching pursuit to raw data. The estimated parameters are mapped to form a SAR image, and the mapping procedure can be implemented under application guidelines. This algorithm requires no prior information about the relative motion between the platform and the target. The Cramer-Rao bounds of parameter estimation are derived, and the root mean square errors of the estimates are close to the bounds. Experimental results are given to validate the algorithm and indicate its potential applications.
Study on Superpixel-Level Sea Clutter Statistical Model for SAR Imagery

Abstract:With the development of remote sensing technology, the acquired SAR images are gradually developing toward high resolution and large scale. At the same time, the interpretation of remote sensing images has also evolved from the traditional pixel-based processing method to the object-based processing method to meet the need of real-time processing. In this paper, we find that the SciPy statistical function library (SPSFL) can provide more matched distribution models for sea clutters than traditionally used models through experiments on SAR images. Thus, we innovatively using the SPSFL to analyze the distribution model of superpixel-level sea clutters, and the experiment results indicate that the Johnsonsu distribution model fits the superpixel-level sea clutters best under different conditions. In addition, this conclusion is verified by multiple sets of experiments. Research results of this paper can provide theoretical and experimental support for the sea clutters distribution models in superpixel-level remote sensing image interpretation.
SAR Image Segmentation Based on Multiscale AutoRegressive and Markov Random Field Models

Abstract:A method of SAR image segmentation based on Multiscale AutoRegressive and Markov Random Field (MAR-MRF) models is presented. MAR models is used to establish mathematic relationship among different image layers, and is combined with Markov Random Field (MRF) segment models. This method takes into account the dependence of neighbor layers Markov property of the same layer, and uses forecasting result of the MAR models to direct the fine layer segmentation. Experimental results on SAR image show that this method reduces the iterative times of segmentation and inaccuracy classify blocks, and gets clear and smooth object border.

Abstract:© 2019 IEEE. This article proposes a generalized modeling and simulation approach for correlated synthetic aperture radar (SAR) texture based on the Gaussian coherent scatterer model. It is rooted in the physics-based coherent scatterer assumption where each observation in an SAR image is a coherent sum of multiple underlying Gaussian scatterers. The proposal generalizes existing single-point statistical models by allowing the number of scatterers to be a correlated random field. It can also generate the desired spatial correlation texture by stipulating the structure in both the Gaussian scattered field and the number of scatterers. This generalized model is derived theoretically and then validated by both simulations and experiments with SAR data from actual sensors.
