Abstract:The real-time prediction of tunnel boring machine (TBM) driving parameters is a critical step during the process of tunnel excavation. The experimental results for TransTP promise superiority, which achieves a state-of-the-art performance for the TBM driving parameter prediction dataset.

Abstract:This paper investigates the prediction of geological conditions ahead of tunnel boring machines (TBM) using a hybrid deep learning approach. By integrating graph convolutional network (GCN) and long short-term memory (LSTM) networks, the spatial and temporal features from TBM parameters and geological information are extracted for accurate prediction. The results from the case study indicate that (1) The proposed approach provides estimation with a high accuracy of 0.9986; (2) The past geological information has a significant contribution to the model; (3) The proposed approach outperforms several state-of-the-art methods including support vector machine (SVM), extreme gradient boosting (XGBoost) and LSTM method. The proposed hybrid deep learning approach can be a useful tool that provides reliable estimation of the advanced geological conditions in real-time.

Abstract:Based on the investigation and analysis of the traffic volume in highway tunnel group region, the development trend of traffic volume is analyzed by Grey model. Then the prediction accuracy is improved by Markov optimization. The method in this paper has a better prediction accuracy and practicality in a period than other common prediction methods. It can be used for the prediction analysis of traffic volume and for early warning by highway management.

Abstract:Rockburst is a common engineering geological disaster in deep rock excavations.To evaluate the possibility of rockburst,a rockburst prediction method using the particle swarm optimization(PSO) algorithm and the general regression neural network(GRNN) model is proposed.This approach employs the technology of neural network to build up a regression model based on existing rockburst database,and takes advantage of PSO algorithm to optimize the parameters of the network which is believed to reduce the adverse influence of man-induced factors in model construction.Then,four major influence factors,including the maximum induced tangential stress on the boundaries of tunnels or caverns,the uniaxial compressive strength and the uniaxial tensile strength of the rock,and also the elastic energy index of the rock,are selected as the inputs for establishing the PSO-GRNN model based on the energy theory and the data obtained from 26 practical cases.The generated PSO-GRNN model is finally applied to predict the rockburst for the Cangling tunnel and Dongguashan copper mine,in which the feasibility and applicability of the proposed approach are illustrated.The methodology presented in the paper provides a reference for some similar engineering involving rockburst.

Abstract:Urban subway tunnel construction inevitably disturbs the surrounding rock and causes the deformation of existing subway structures. Dynamic predictions of the tunnel horizontal displacement, tunnel ballast settlement, and tunnel differential settlement are important for ensuring the safety of buildings and tunnels. First, based on the Hangzhou Metro project, we analyzed the influence of construction on the deformation of existing subway structures and the difficulties and key points in monitoring. Then, a deformation prediction model, based on a back propagation (BP) neural network, was established with massive monitoring data. In particular, we analyzed the influence of four structures of the BP neural network on prediction performance, i.e., single input-single hidden layer–single output, multiple inputs–single hidden layer–single output, single input–double hidden layers–single output, and multiple inputs–double hidden layers-single output, and verified them using measured data.

Abstract:Tunnel boring machine (TBM) is a complex engineering system widely used for tunnel construction. In view of the complicated construction environments, it is necessary to predict geology conditions prior to excavation. In recent years, massive operation data of TBM has been recorded, and mining these data can provide important references and useful information for designers and operators of TBM. In this work, a geology prediction approach is proposed based on deep neural network and operation data. It can provide relatively accurate geology prediction results ahead of the tunnel face compared with the other prediction models based on statistical learning methods. The application case study on a tunnel in China shows that the proposed approach can accurately estimate the geological conditions prior to excavation, especially for the short range ahead of training data. This work can be regarded as a good complement to the geophysical prospecting approach during the construction of tunnels, and also highlights the applicability and potential of deep neural networks for other data mining tasks of TBMs.
Dynamic prediction for attitude and position of shield machine in tunneling: A hybrid deep learning method considering dual attention

Abstract:In constructing long-distance shield tunnels, it is a difficult challenge to maintain the tunneling trajectory consistent with the design tunnel axis. The accurate prediction of the attitude and position during tunneling can reap the advantage of optimizing the tunneling operation parameters in advance leading to the best tunneling trajectory. This study investigates a framework based on a hybrid deep learning model for attitude and position prediction of the shield machine. This prediction framework contains comprehensive feature evaluation method, ensemble empirical mode decomposition (EEMD), convolutional neural network (CNN), and gate recurrent unit (GRU). The introduction of channel attention and temporal attention in CNN and GRU further strengthens the spatial and temporal feature extraction ability of the model. The performance of the prediction framework is verified through a case study with data collected from the Shanghai urban railway tunnel section. Results reveal that the proposed model with dual attention significantly outperforms other models in prediction accuracy and speed. The bias of feature data can be alleviated by introducing channel attention, and using temporal attention can capture long-distance temporal feature data. The model can support shield construction safety by adjusting the operation parameters, and an application example is used to demonstrate the feasibility of the proposed approach.

Abstract:This study proposes a hybrid deep learning approach for dynamic attitude and position prediction of the tunnel boring machine (TBM) with high accuracy. By utilizing the key operational parameters as well as the historical value of TBM’s positions, the proposed deep learning model with graph convolutional network (GCN) and long short-term memory (LSTM), named GCN-LSTM, is constructed and trained to predict the vertical and horizontal deviations at the articulation and tail of TBM. Shapley Additive exPlanations (SHAP) analysis is then performed to improve the model’s interpretability and determine the key contributing factors. Data obtained from a realistic tunnel project in Singapore’s Thomson-East Coast line is utilized as a case study. The results indicate that: (1) The proposed GCN-LSTM approach provides accurate prediction with an average MAE of 1.009 mm, RMSE of 1.445 mm and R2 of 0.941. (2) The historical values of the deviation and adjustment are the major contributions to the current deviations, while the present adjustment could only influence the deviation in the future. (3) The proposed GCN-LSTM model outperforms the state-of-the-art methods in most metrics for the four outputs and thus is the most suitable method for the prediction. The proposed approach provides a reliable estimation of TBM’s position which assists in improving the overall project quality and reduces the risk of tunnel misalignments.

Predicting the Performance of Tunnel Boring Machines using Big Operational Data

Abstract:Accurate prediction of the performance of tunnel boring machines (TBMs) is important to safe and efficient tunneling. Traditional prediction method of TBM performance is restricted by the lack of sufficient rock mass data and the prediction accuracy is low. A comprehensive management and preprocessing framework of TBM big operational data is proposed in this paper, after which a new prediction method of TBM performance is proposed. The effectiveness of the proposed method is tested on 4 different tunnels. Prediction results show that the big operational data based method can predict TBM performance with high accuracy, and in most cases, the random forest algorithm generates better prediction results than the long-short term memory (LSTM) neural network. The data imbalance phenomenon leads to the emergence of big prediction errors on certain operational segments, highlighting the necessity of adopting new sampling methods to create a more balanced dataset, and incremental learning methods to update the prediction model timely.

Abstract:One main challenge in tunnel constructions is to predict the tunnel geological conditions without excavation to ensure safety during the construction process. This paper proposes a data-driven framework for real-time interpreting the operating data of tunnel boring machines (TBMs) without interrupting tunneling operations, and eventually automate the tunneling operation. In this framework, we first convert the indexes of the original data from discontinuous operating time to continuous operating displacement. After screening outliers, to more exhaustively explore the inherent characteristics of the TBM operating data, we then augment features by using the first-order and the second-order difference information. There are two main concerns for developing a desired geological-type predictor: 1) since multiple geological types could coexist in one tunnel section, the predictor should have multiple outputs and 2) since the geological types are specified by the values of 7 kinds of physical-mechanical indexes of geological types, this geological characteristic should also be encoded into the predictor’s structure. Therefore, we design a feed-forward multiple-output artificial neural network (ANN) with two hidden layers as the predictor, where the second hidden layer has 7 nodes that correspond to 7 kinds of physical-mechanical indexes. The experimental results show that: 1) the feature augmentation (FA) method indeed improves the prediction performance; 2) the ANN predictor has the best performance on the test set when the second hidden layer has 7 nodes; 3) the proposed ANN predictor outperforms many widely-used learning models, e.g., XGboost, random forest (RF), and support vector regression (SVR); and 4) the predictor is capable of accurately predicting the geological types of stratum.

Abstract:A tunnel boring machine (TBM) is a type of heavy load equipment that is widely used in underground tunnel construction. The geological conditions in the tunneling process are decisive factors that directly affect the control of construction equipment. Because TBM tunneling always takes place underground, the acquisition of geological information has become a key issue in this field. This study focused on the internal relationships between the sequential nature of tunnel in situ data and the continuous interaction between equipment and geology and introduced the long short-term memory (LSTM) time series neural network method for processing in situ data. A method for predicting the geological parameters in advance based on TBM real-time state monitoring data is proposed. The proposed method was applied to a tunnel project in China, and the R2 of the prediction results for five geological parameters are all higher than 0.98. The performance of the LSTM was compared with that of an artificial neural network (ANN). The prediction accuracy of the LSTM was significantly higher compared with that of the ANN, and the generalization and robustness of LSTM are also better than those of ANN, which indicates that the proposed LSTM method could extract the sequence properties of the in situ data. The rule of equipment-geology interaction was reflected by increasing the memory structure of the model through the introduction of the “gate” concept, and the accurate prediction of geological parameters during tunneling was realized. Additionally, the influence of time window and distance of prediction on the model is discussed. The proposed method provides a new approach toward obtaining geological information during TBM construction and also provides a certain reference for the effective analysis of the in situ data with sequence properties.

Abstract:This work explores the potential for predicting TBM performance using deep learning. It focuses on a 17.5-km-long tunnel excavated for the Yingsong Water Diversion Project in Northeastern China with its 728 days' continuous monitoring of mechanical data. The prediction uses the deep belief network (DBN) proposed by Hinton et al. (2006),on the penetration rate, cutter rotation speed, torque, and thrust force. Field Penetration Index (FPI) is introduced to quantify TBM performance in the field. The DBN algorithm trains on nth number of preceding elements and predicts the performance of the n + 1th element. Prior to the implementation of the DBN, a pilot test was performed to find the optimal values for the network structural parameters (number of input nodes, number of hidden layers, number of nodes in the hidden layers, and learning rate). Predictions on FPIs in all the three rock types were then proceeded with good agreement with the field measured data. The mean relative errors for the predicted measured FPIs are generally less than 0.15 and the correlation coefficients (R) can be higher than 0.78. The predicted and measured FPI values along the length of the tunnel graphically follow the same trends. These results confirm the usefulness of big data and the deep learning in predicting TBM performance.
Tunnel deformation prediction during construction: An explainable hybrid model considering temporal and static factors

Abstract:This paper presents a novel hybrid model designed for predicting mountain tunnel deformation during construction, incorporating both temporal and static factors. Utilizing a boosting ensemble technique, the model effectively integrates a bidirectional Long Short-Term Memory (Bi-LSTM) network—acclaimed for its proficiency with time-series data—with the Light Gradient Boosting Machine (Light GBM) model—recognized for its adept handling of tabular data. In the prediction procedure, the Bi-LSTM and Light GBM modules are engaged to process time-dependent and static factors, respectively. The model's performance was evaluated against seven other established machine learning models using data from the Liangwangshan Tunnel, whose outcomes demonstrated the superiority of our model in terms of its local and overall reduction in prediction errors. By introducing static factors associated with each monitoring section via the Light GBM, our model offers a robust solution to the issue of time delayed prediction—a challenge inadequately addressed in time series prediction. Finally, we used the SHAP (SHapley Additive exPlanations) method to interpret the hybrid model's decision-making mechanisms. The findings reveal a significant correlation between the prediction rules employed by our model and the fundamental principles of tunnel engineering and physical mechanics, thereby underlining its reliability and potential applicability in practical scenarios.

Abstract:This study presents a hybrid model based on the particle swarm optimization (PSO) algorithm and a long shortterm memory (LSTM) neural network. PSO can determine the hyperparameters for the LSTM neural network. Using this approach, a framework for automatic data collection and application of the developed model during tunnel excavation was explored. The proposed model includes three stages: (i) data collection and preprocessing, (ii) hybrid prediction model establishment, and (iii) model performance validation. Pearson correlation coefficient is adopted to analyze the relationships between the influential factors and predicted object, which aids in feature selection for the developed model. A total of 1500 data sets, from a tunnel construction case in Shenzhen, China, were collected for training and testing the hybrid model. The results showed that the hybrid model with all the influential factors yielded the best performance. Thus, the developed model can provide a guideline for coping with measured data from an automatic monitoring system in earth pressure balance shield machines.

Abstract:Displacement prediction of tunnel surrounding rock plays an important role in safety monitoring and quality control tunnel construction. In this paper, two methodologies, support vector machines (SVM) and artificial neural network (ANN), are introduced to predict tunnel surrounding rock displacement. Then the two modes are texted with the data of Fangtianchong tunnel, respectively. The comparative results show that solutions gained by SVM seem to be more robust with a smaller standard error compared to ANN. Generally, the comparison between artificial neural network (ANN) and SVM shows that SVM has a higher accuracy prediction than ANN. Results also show that SVM seems to be a powerful tool for tunnel surrounding rock displacement prediction.

Abstract:Accurately predicting tunnel boring machine (TBM) performance is beneficial for excavation efficiency enhancement and risk mitigation of TBM tunneling. In this paper, we develop a long short-term memory (LSTM) based hybrid intelligent model to predict two key TBM performance parameters (advance rate and cutterhead torque). The model combines the LSTM, BN, Dropout and Dense layers to process the raw data and improve the fitting quality. The features, including the ground formation properties, tunnel route curvature, tunnel location and TBM operational parameters, are divided into historical/real-time time-varying parameters, time-invariant parameters and historical/real-time output prediction data. The effectiveness of the proposed model is verified based on a large monitoring database of the Baimang River Tunnel Project in Shenzhen, south China. We then discuss the influence of the prediction mode, neural network structure and time division interval length of historical data on the prediction accuracy. The significance evaluation of input features shows that the historical output prediction has the largest influence on the prediction accuracy, and the influence of ground properties is secondary. It is also found that the correlations between input features and the output prediction are coincident with their interrelationships with the ground properties and ease of TBM excavation. Finally, it is found that the prediction results are most affected by the total propulsion force followed by the rotation speed of the cutterhead. The established model can provide useful guidance for construction personnel to roughly grasp the possible TBM status from the prediction results when adjusting the operational parameters.

Abstract:Accurate prediction of the future mechanical behaviour of the underground structure is important for the traffic system. However, the existing works mostly just predicted one type of property and failed to study the influence of different properties in the tunnel. Besides, most of them predicted future behaviours without considering the external influence of the environment like temperature and water pressure. In this paper, we propose a multi-task prediction model named MSTNet which combines different types of indicators and external factors for capturing the temporal and spatial characteristics in the tunnel. Firstly, we integrate time series of multiple indicators and build a deep learning algorithm based on a graph neural network and recurrent network to capture the temporal, spatial and external impacts in the tunnel. Then, we have a case study on the Wuhan Yangtze River tunnel which contains the comparison of different components in our model, the compared results between the single indicator and multiple indicators and the performance analysis among traditional models. From the experiment results, we could find that the ability of the MSTNet model is superior to other methods, whose capability achieved over 93% and 94% in strain variation and joint opening sensors on Pearson Correlation Coefficient (PCC) in the next 45 days, respectively.

Abstract:Accurately predicting the performance of a tunnel boring machine (TBM) is important to safe and efficient tunneling. The application of machine learning algorithms to TBM performance prediction creates several challenges. Such prediction is a nontrivial task involving procedures such as data preprocessing, selection of a machine learning algorithm and optimization of the related hyperparameters. The demand for expert knowledge has restricted the application of machine learning methods to TBM performance prediction, and it is meaningful to study predicting TBM performance automatically. In this paper, we explore three approaches to TBM performance prediction using Bayesian optimization and automated machine learning (AutoML). In the first study, Bayesian optimization is used to determine the optimal hyperparameters of various machine learning algorithms, including support vector regression (SVR), decision tree, bagging tree, random forest and AdaBoost. We attain the minimum mean squared error (MSE) values of 3.135 x 10(-2) and 3.177 x 10(-2) for a decision tree and SVR, respectively. In the second approach called the neural architecture search (NAS), the optimal combination of architecture, hyperparameters and the training procedure of an artificial neural network is found in a single operation. We obtain the optimal results of 3.514 x 10(-2) and 3.237 x 10(-2) if complete and simplified NAS are used, respectively. In the third method, the best combination of a data preprocessing method, a machine learning model and the related hyperparameters is found, and an optimal MSE value of 3.148 x 10(-2) is obtained using AutoML. In all three studies, we obtain state-of-the-art prediction results that are superior to a previous best prediction result of 3.500 x 10(-2). The prediction results prove that Bayesian optimization and AutoML are powerful tools that can not only effectively predict TBM performance but also reduce the demand for expert knowledge of machine learning.

Abstract:This paper presents a comprehensive procedure to predict geological conditions (i.e., rock mass types) for a tunneling boring machine (TBM) based on big operational data including four channels: cutterhead speed, cutterhead torque, thrust, and advance rate. To handle the big operational data, a Balanced Iterative Reducing and Clustering using Hierarchies (BIRCH) algorithm is adopted to effectively compress 12,038,636 TBM operational data to only 5014 leaf node entries. A K-means++ algorithm is used to find potential rock mass types in the TBM operational data. By comparing three kinds of classifiers, a support vector classifier (SVC) with an average precision of 98.6% is selected as the best geological conditions prediction model. Test results on historical TBM operational segments show that most adjacent operational segments have the same rock mass type. The change in rock mass type is a dynamic process, which first fluctuates between two rock mass types and gradually stabilizes at the latter type. In addition, the cutterhead torque and thrust are found to better reflect the change of rock mass types compared with the advance rate and cutterhead speed. Test results on a water conveyance tunnel show that using only 20% of TBM training data the developed prediction model can generate 84.4% precision and 88.8% recall performance for the remaining 80% testing data. Hence, the proposed procedure could be applied to big TBM operational data to accurately detect, characterize, and predict rock mass types, which is of critical importance to safe and efficient tunneling.
