Abstract:With the rapid development of the Internet and the approaching of the next-generation networking, the number and variety of delay-sensitive applications have increased dramatically. Nowadays, how to properly route delay-sensitive packets in complex network environment and meet the stringent quality-of-service (QoS) requirements of delay-sensitive applications remains a great challenge. Towards this end, this paper proposes a deep reinforcement learning (DRL)-based routing algorithm for delay-sensitive applications featuring the proximal policy optimization (PPO) method and the front-convergent actor-critic network (FCACN) technique. To meet the high demand of delay-sensitive applications, we consider the packet survival time (ST) to help our algorithm perform better and make up for the shortage of the time-to-live (TTL) mechanism in IP network. We conduct extensive experiments to prove the efficiency and reliability of the proposed algorithm. Experimental results show that the proposed algorithm outperforms two traditional routing protocols and two state-of-the-art DRL-based routing algorithms in terms of minimizing delay and packet loss rate.

Abstract:Traditional routing algorithms cannot dynamically change network environments due to the limited information for routing decisions. Meanwhile, they are prone to performance bottlenecks in the face of increasingly complex business requirements. Some approaches, such as deep reinforcement learning (DRL) have been proposed to address the routing problems. However, they hardly utilize the information about the network environment fully. The Knowledge Defined Networking (KDN) architecture inspires us to develop new learning mechanisms adapted to the dynamic characteristics of the network topology. In this paper, we propose an effective scheme to solve the routing optimization problem by adding a graph neural network (GNN) structure to DRL, called Message Passing Deep Reinforcement Learning (MPDRL). MPDRL uses the characteristics of GNN to interact with the network topology environment and extracts exploitable knowledge through the message passing process of information between links in the topology. The goal is to achieve the load balance of network traffic and improve network performance. We have conducted experiments on three Internet Service Provider (ISP) network topologies. The evaluation results show that MPDRL obtains better network performance than the baseline algorithms.

Towards Cognitive Routing based on Deep Reinforcement Learning

Abstract:Routing is one of the key functions for stable operation of network infrastructure. Nowadays, the rapid growth of network traffic volume and changing of service requirements call for more intelligent routing methods than before. Towards this end, we propose a definition of cognitive routing and an implementation approach based on Deep Reinforcement Learning (DRL). To facilitate the research of DRL-based cognitive routing, we introduce a simulator named RL4Net for DRL-based routing algorithm development and simulation. Then, we design and implement a DDPG-based routing algorithm. The simulation results on an example network topology show that the DDPG-based routing algorithm achieves better performance than OSPF and random weight algorithms. It demonstrate the preliminary feasibility and potential advantage of cognitive routing for future network.

A Routing Optimization Method for Software-Defined SGIN Based on Deep Reinforcement Learning

Abstract:As space networks become more and more important, the Space-ground Integration network (SGIN) has received unprecedented attention. However, dynamic changes of topology and link status of satellite networks bring many challenges to routing optimization in the SGIN. Traditional routing optimization methods do not perform well, as they do not consider changes of topology and link status, as well as the association between flows. Since the Machine Learning (ML) technologies have shown significant advantages in dynamic routing optimization, we proposed a Machine Learning-based Space-ground Integration Networking (ML-SSGIN) framework that combines Software-Defined Networking (SDN) technologies to solve this challenge. To evaluate the feasibility of the proposed framework, the Deep Deterministic Policy Gradient (DDPG), a Deep Reinforcement Learning (DRL) algorithm, is deployed to perform routing optimization, which can make routing decisions based on real-time link status. In particular, we utilize a neural network that integrates Long Short-Term Memory Network (LSTM) and Dense layers for its actor and critic part to improve perceptual capabilities of contextual correlations between flows. We compared the proposed DDPG neural network with the one only having the Dense layers. The results show that the proposed architecture is feasible and effective. What's more, compared to Open Shortest Path First (OSPF) algorithm, our proposed routing optimization method can adapt to continuously change flows, and link status, which improves end-to-end throughput and latency.

Abstract:Routing optimization has long been a problem in the networking field. With the rapid development of user applications, network traffic is continuously increasing in dynamicity, making optimization of the routing problem NP-hard. Traditional routing algorithms cannot ensure both accuracy and efficiency. Deep reinforcement learning (DRL) has recently shown great potential in solving networking problems. However, existing DRL-based routing solutions cannot process the graph-like information in the network topology and do not generalize well when the topology changes. In this paper, we propose AutoGNN, which combines a GNN and DRL for the automatic generation of routing policies. In AutoGNN, the traffic distribution in the network topology is processed by a GNN, while a DRL framework is used to train the parameters of neural networks without human expertise. Our experimental results show that AutoGNN can improve the average end-to-end delay of the network by up to 19.7% as well as present more robustness against topology changes.

Abstract:Due to the highly dynamic changes in wireless network topologies, efficiently obtaining network status information and flexibly forwarding data to improve communication quality of service are important challenges. This article introduces an intelligent routing algorithm (DRL-PPONSA) based on proximal policy optimization deep reinforcement learning with network situational awareness under a software-defined wireless networking architecture. First, a specific data plane is designed for network topology construction and data forwarding. The control plane collects network traffic information, sends flow tables, and uses a GCN-GRU prediction mechanism to perceive future traffic change trends to achieve network situational awareness. Second, a DRL-based data forwarding mechanism is designed in the knowledge plane. The predicted network traffic matrix and topology information matrix are treated as the environment for DRL agents, while next-hop adjacent nodes are treated as executable actions. Accordingly, action selection strategies are designed for different network conditions to achieve more intelligent, flexible, and efficient routing control. The reward function is designed using network link information and various reward and penalty mechanisms. Additionally, importance sampling and gradient clipping techniques are employed during gradient updating to enhance convergence speed and stability. Experimental results show that DRL-PPONSA outperforms traditional routing methods in network throughput, delay, packet loss rate, and wireless node distance. Compared to value-function-based Dueling DQN routing, the convergence speed is significantly improved, and the convergence effect is more stable. Simultaneously, its consumption of hardware storage space is reduced, and efficient routing decisions can be made in real-time using the current network state information.

Abstract:To enhance the efficiency and expediency of issuing e-licenses within the power sector, we must confront the challenge of managing the surging demand for data traffic. Within this realm, the network imposes stringent Quality of Service (QoS) requirements, revealing the inadequacies of traditional routing allocation mechanisms in accommodating such extensive data flows. In response to the imperative of handling a substantial influx of data requests promptly and alleviating the constraints of existing technologies and network congestion, we present an architecture for QoS routing optimization with in Software Defined Network (SDN), leveraging deep reinforcement learning. This innovative approach entails the separation of SDN control and transmission functionalities, centralizing control over data forwarding while integrating deep reinforcement learning for informed routing decisions. By factoring in considerations such as delay, bandwidth, jitter rate, and packet loss rate, we design a reward function to guide the Deep Deterministic Policy Gradient (DDPG) algorithm in learning the optimal routing strategy to furnish superior QoS provision. In our empirical investigations, we juxtapose the performance of Deep Reinforcement Learning (DRL) against that of Shortest Path (SP) algorithms in terms of data packet transmission delay. The experimental simulation results show that our proposed algorithm has significant efficacy in reducing network delay and improving the overall transmission efficiency, which is superior to the traditional methods.

Abstract:The rapid development of wireless communications brings a tremendous increase in the amount number of data streams and poses significant challenges to the traditional routing protocols. In this paper, we leverage deep reinforcement learning (DRL) for router selection in the network with heavy traffic, aiming at reducing the network congestion and the length of the data transmission path. We first illustrate the challenges of the existing routing protocols when the amount of the data explodes. We then utilize the Markov decision process (RSMDP) to formulate the routing problem. Two novel deep Q network (DQN)-based algorithms are designed to reduce the network congestion probability with a short transmission path: one focusing on reducing the congestion probability; while the other focuses on shortening the transmission path. The simulation results demonstrate that the proposed algorithms can achieve higher network throughput comparing to existing routing algorithms in heavy network traffic scenarios.

Abstract:Mobile Edge Computing (MEC) has solved a sharp increase in data volume caused by various emerging network applications. The edge data center is an essential part of MEC, which connects the edge of the network and the backbone network. Faced with a complex network environment, edge data centers suffer low bandwidth resource utilization and high network latency. This paper proposes Twin Delayed Deep Deterministic policy gradient based Routing Optimization (TRO) algorithm to improve the performance of edge data centers. The TRO algorithm uses Deep Reinforcement Learning (DRL) and Software-Defined Networking (SDN) to achieve routing optimization from two aspects of bandwidth utilization and load balancing. Experiments demonstrate that compared with other algorithms, the TRO algorithm proposed in this paper significantly improves network throughput and reduces average packet latency and average packet latency error.
Adaptive and Robust Network Routing Based on Deep Reinforcement Learning with Lyapunov Optimization.

Abstract:The most recent development of the Internet of Things brings massive timely-sensitive and yet bursty data flows. The adaptive network control has been explored using deep reinforcement learning, but it is not sufficient for extremely bursty network traffic flows, especially when the network traffic pattern may change over time. We model the routing control in an environment with time-variant link delays as a Lyapunov optimization problem. We identify that there is a tradeoff between optimization performance and modeling accuracy when the propagation delays are included. We propose a novel deep reinforcement learning-based adaptive network routing method to tackle the issues mentioned above. A Lyapunov optimization technique is used to reduce the upper bound of the Lyapunov drift, which leads to improved queuing stability in networked systems. Experiment results show that the proposed method can learn a routing control policy and adapt to the changing environment. The proposed method outperforms the baseline backpressure method in multiple settings, and converges faster than existing methods. Moreover, the deep reinforcement learning module can effectively learn a better estimation of the long-term Lyapunov drift and penalty functions, and thus it provides superior results in terms of the backlog size, end-to-end latency, age of information, and throughput. Extensive experiments also show that the proposed model performs well under various topologies, and thus the proposed model can be used in general cases. Also the user can adjust the preference parameter at ant time without the need to retrain the neural networks.
Improving the Scalability of Deep Reinforcement Learning-Based Routing with Control on Partial Nodes

Abstract:Machine Learning (ML)-based routing optimization has been proposed to optimize the performance of flow routing for future networks, such as Software-Defined Networks (SDNs). However, existing studies are either hard to converge for large networks or vulnerable to topology changes. In this paper, we propose SINET, a scalable and intelligent network control framework for routing optimization. To improve the robustness and scalability, SINET selects several critical routing nodes to be directly controlled by a Deep Reinforcement Learning (DRL) agent, which dynamically generates routing policy to optimize network performance. Simulation results show that SINET can reduce the average flow completion time by at least 32% for a network with 82 nodes and exhibit better robustness against minor topology changes, compared to other DRL-based schemes.

Abstract:With the continuous development of network technologies such as cloud computing and mobile computing, the demand of services is increasing significantly, which brings exponential grow of network traffic. In order to solve the routing problem of high concurrent traffic on the premise of ensuring QoS, an intelligent routing optimization mechanism is needed to realize the traffic efficient forwarding. Software-defined networks(SDN) provide the basis for programmable routing. Additionally, SDN and IPv6 are compatible with natural programmable capabilities, and technologies such as BIERv6 and iFIT can be deployed on it. In SDN, the controller can control the traffic routing by modifying the routing table in the switch, but the inefficient routing decision will lead to the overload of the network link and increase the end-to-end transmission delay. Deep reinforcement learning has the ability of intelligent decision-making and processing large-scale high-dimensional data, which is suitable for solving decision optimization problems such as network routing decision-making. In this paper, we proposed an intelligent routing optimization model based on SDN. The model uses deep reinforcement learning to learn the relationship between the traffic load of switches and network performance, and uses Nadam optimizer to update gradients to determine the link weights in the network. SDN controller determines the routing forwarding path through the link weights.
Packet Routing Against Network Congestion: A Deep Multi-agent Reinforcement Learning Approach

Abstract:The continuous growth of the network data would lead to the increased network congestion and the throughput decline. In this paper, we investigate the packet routing problem based on deep multi-agent reinforcement learning, where each router chooses the next hop router by itself intelligently. We design the modified deep Q-network in each router to evaluate the neighbor routers. The routers, each acting as an agent, choose the next hop router based on their local observation. Then they transfer the packets to the chosen routers and receive the reward and the observation of the next hop routers. Using their experience, the routers learn to improve the packet routing strategy by updating their Q-networks. We demonstrate that with proper reward set and training mechanism, the routers in the network can work in a distributed way to reduce the computational complexity compared with the single-agent reinforcement learning based algorithm. And the proposed algorithm can further reduce the congestion probability and improve the network performance.

Abstract:Wireless sensor network is a network that integrates sensor technology, computer technology, information processing technology, and communication technology. This paper aims to study how to analyze and study the routing optimization of wireless sensor network based on deep learning and describe the neural network. This paper puts forward the problem of routing optimization, which is based on the dynamic programming of wireless sensor network, and then elaborates around its concept and related algorithms and designs and analyzes the case of wireless sensor network optimization. Through the comparative analysis of the five algorithms in computer simulation, although the average network delay performance of DPER reached 0.47 s, it could effectively prolong the life cycle of the network. The DPER algorithm not only improves the network life but also improves the network energy utilization rate, shortens the average path length of the network, and reduces the standard deviation of the remaining energy of the node.

Abstract:This paper proposes DROM, a deep reinforcement learning mechanism for Software-Defined Networks (SDN) to achieve a universal and customizable routing optimization. DROM simplifies the network operation and maintenance by improving the network performance, such as delay and throughput, with a black-box optimization in continuous time. We evaluate the DROM with experiments. The experimental results show that DROM has the good convergence and effectiveness and provides better routing configurations than existing solutions to improve the network performance, such as reducing the delay and improving the throughput.
A Hybrid Deep Reinforcement Learning Routing Method under Dynamic and Complex Traffic with Software Defined Networking

Abstract:Software-defined networking (SDN) routing based on reinforcement learning (RL) is a very promising research topic in recent years, achieving better solutions comparing to traditional network routing based on mathematical models. However, with continuous increase of network complexity and scale, the RL methods show a slow convergence speed and insufficient adaptability to network changes. This leads to the major drawbacks of existing RL algorithms in modern large-scale networks, especially with complexity and dynamics features. Therefore, this paper proposed a novel RL method based on pre-trained data called PRLR, a pre-trained reinforcement learning based SDN routing method, which can effectively improve the QoS of SDN routing and improve the convergence speed of reinforcement learning. The experimental results demonstrate that our proposed PRLR outperforms the benchmarking methods in terms of multiple metrics, such as network delays, bandwidth availability, goodput ratio, as well as the convergence efficiency and works well in dynamic routing topologies.
Deep Distributional Reinforcement Learning-Based Adaptive Routing with Guaranteed Delay Bounds

Abstract:Real-time applications that require timely data delivery over wireless multi-hop networks within specified deadlines are growing increasingly. Effective routing protocols that can guarantee real-time QoS are crucial, yet challenging, due to the unpredictable variations in end-to-end delay caused by unreliable wireless channels. In such conditions, the upper bound on the end-to-end delay, i.e., worst-case end-to-end delay, should be guaranteed within the deadline. However, existing routing protocols with guaranteed delay bounds cannot strictly guarantee real-time QoS because they assume that the worst-case end-to-end delay is known and ignore the impact of routing policies on the worst-case end-to-end delay determination. In this paper, we relax this assumption and propose DDRL-ARGB, an Adaptive Routing with Guaranteed delay Bounds using Deep Distributional Reinforcement Learning (DDRL). DDRL-ARGB adopts DDRL to jointly determine the worst-case end-to-end delay and learn routing policies. To accurately determine worst-case end-to-end delay, DDRL-ARGB employs a quantile regression deep Q-network to learn the end-to-end delay cumulative distribution. To guarantee real-time QoS, DDRL-ARGB optimizes routing decisions under the constraint of worst-case end-to-end delay within the deadline. To improve traffic congestion, DDRL-ARGB considers the network congestion status when making routing decisions. Extensive results show that DDRL-ARGB can accurately calculate worst-case end-to-end delay, and can strictly guarantee real-time QoS under a small tolerant violation probability against two state-of-the-art routing protocols.

Abstract:Routing algorithms, which determine how to deliver traffic from the source to the destination, are essential for next-generation networks and the internet. To make optimal routing decisions in complex network environments, researchers have leveraged Deep Reinforcement Learning (DRL) to design next-generation routing mechanisms. However, most existing DRL-based routing algorithms are implemented using traditional Neural Networks (NN), which lack robustness against topology changes. In this paper, we propose a novel algorithm called GAPPO, which integrates Graph Attention Network (GAT) and Proximal Policy Optimization (PPO) to optimize routing policies with the objective of minimizing end-to-end (E2E) latency in networks affected by link failures. To evaluate the performance of the proposed algorithm, we conduct a series of experiments on dynamically changing topologies with link failures under different loads. Experimental results demonstrate that GAPPO outperforms benchmark algorithms in both simulated and real-world networks, confirming its powerful robustness against link failures.

Abstract:Global routing has been a historically challenging problem in electronic circuit design, where the challenge is to connect a large and arbitrary number of circuit components with wires without violating the design rules for the printed circuit boards or integrated circuits. Similar routing problems also exist in the design of complex hydraulic systems, pipe systems and logistic networks. Existing solutions typically consist of greedy algorithms and hard-coded heuristics. As such, existing approaches suffer from a lack of model flexibility and non-optimum solutions. As an alternative approach, this work presents a deep reinforcement learning method for solving the global routing problem in a simulated environment. At the heart of the proposed method is deep reinforcement learning that enables an agent to produce an optimal policy for routing based on the variety of problems it is presented with leveraging the conjoint optimization mechanism of deep reinforcement learning. Conjoint optimization mechanism is explained and demonstrated in details; the best network structure and the parameters of the learned model are explored. Based on the fine-tuned model, routing solutions and rewards are presented and analyzed. The results indicate that the approach can outperform the benchmark method of a sequential A* method, suggesting a promising potential for deep reinforcement learning for global routing and other routing or path planning problems in general. Another major contribution of this work is the development of a global routing problem sets generator with the ability to generate parameterized global routing problem sets with different size and constraints, enabling evaluation of different routing algorithms and the generation of training datasets for future data-driven routing approaches.
