Abstract:We study the problem of approximate nearest neighbor search in $d$-dimensional Hamming space {0,1} d . We study the complexity of the problem in the famous cell-probe model, a classic model for data structures. We consider algorithms in the cell-probe model with limited adaptivity, where the algorithm makes k rounds of parallel accesses to the data structure for a given k. For any k ≥ 1, we give a simple randomized algorithm solving the approximate nearest neighbor search using k rounds of parallel memory accesses, with O(k(log d) 1/k ) accesses in total. We also give a more sophisticated randomized algorithm using O(k+(1/k log d) O(1/k) ) memory accesses in k rounds for large enough k. Both algorithms use data structures of size polynomial in n, the number of points in the database. We prove an Ω(1/k(log d) 1/k ) lower bound for the total number of memory accesses required by any randomized algorithm solving the approximate nearest neighbor search within k ≤ (log log d)/(2 log log log d) rounds of parallel memory accesses on any data structures of polynomial size. This lower bound shows that our first algorithm is asymptotically optimal for any constant round k. And our second algorithm approaches the asymptotically optimal tradeoff between rounds and memory accesses, in a sense that the lower bound of memory accesses for any k 1 rounds can be matched by the algorithm within k 2 =O(k 1 ) rounds. In the extreme, for some large enough k=Θ((log log d)/(log log log d)), our second algorithm matches the Θ((log log d)/(log log log d)) tight bound for fully adaptive algorithms for approximate nearest neighbor search due to Chakrabarti and Regev.

Abstract:The nearest neighbor search is an essential operation for many computer vision, data mining, and machine learning problems. Since it is so widely used, the nearest neighbor search should be as fast as possible. This paper explores lower bound‐based approaches to speed up the exact nearest neighbor search in high dimensional Euclidean space. We compute the lower bound of Euclidean Distance by using the block vectors and Cauchy–Schwartz inequality. The proposed lower bound is calculated efficiently and is close to the real Euclidean Distance. Besides, the preprocessing step of the proposal has linear time complexity. Given a query, during the procedure of identifying the nearest neighbor, our method can eliminate many expensive actual distance computations using the lower bound to approximate Euclidean Distance. In addition, we develop a multilevel lower bound strategy, which calculates the lower bound step by step and utilizes the multistep filtering mechanism to improve the searching process further. Theoretical analysis is provided to show that the proposals can guarantee to obtain the same result as the brute‐force search. Comprehensive experiments on 16 public data sets collected from various domains demonstrate that our approach performs well in finding the exact nearest neighbor compared to related competitors. The experimental results also illustrate that the multilevel lower bound strategy is effective.
Efficient Nearest Neighbor Search in High Dimensional Hamming Space

Abstract:•We address the problem of fast approximate nearest neighbor searching (ANN) in high dimensional Hamming space.•Two existing techniques (LPP and KD-Tree) are combined in a novel and smart manner to achieve an elegant solution of the studied problem, while neither of them is competent for the studied problem.•Detailed analysis on complexity and performance of the proposed method has been supplied.•Extensive experiments with comparison to the state of the art have been reported to validate the effectiveness of the proposed method. The proposed method improves the searching accuracy of the state of the art by 30% (from 60% to 90%) when the searching speed maintains two orders of magnitude faster than the linear scan for a one million database. The speed up factor is even higher for larger database.
An Optimal Randomized Cell Probe Lower Bound for Approximate Nearest Neighbor Searching

Abstract:We consider the approximate nearest neighbor search problem on the Hamming cube $\{0,1\}^d$. We show that a randomized cell probe algorithm that uses polynomial storage and word size $d^{O(1)}$ requires a worst case query time of $\Omega({\rm log}\,{\rm log}\,d/{\rm log}\,{\rm log}\,{\rm log}\,d)$. The approximation factor may be as loose as $2^{{\rm log}^{1-\eta}d}$ for any fixed $\eta>0$. Our result fills a major gap in the study of this problem since all earlier lower bounds either did not allow randomization [A. Chakrabarti et al., A lower bound on the complexity of approximate nearest-neighbor searching on the Hamming cube, in Discrete and Computational Geometry, Springer, Berlin, 2003, pp. 313328; D. Liu, Inform. Process. Lett., 92 (2004), pp. 2329] or did not allow approximation [A. Borodin, R. Ostrovsky, and Y. Rabani, Proceedings of the 31st Annual ACM Symposium on Theory of Computing, 1999, pp. 312321; O. Barkol and Y. Rabani, Proceedings of the 32nd Annual ACM Symposium on Theory of Computing, 2000, pp. 388396; T. S. Jayram et al., J. Comput. System Sci., 69 (2004), pp. 435447]. We also give a cell probe algorithm that proves that our lower bound is optimal. Our proof uses a lower bound on the round complexity of the related communication problem. We show, additionally, that considerations of bit complexity alone cannot prove any nontrivial cell probe lower bound for the problem. This shows that the richness technique [P. B. Miltersen et al., J. Comput. System Sci., 57 (1998), pp. 3749] used in a lot of recent research around this problem would not have helped here. Our proof is based on information theoretic techniques for communication complexity, a theme that has been prominent in recent research [A. Abstract:Approximate K Nearest Neighbor (AKNN) search in high-dimensional spaces is a critical yet challenging problem. In AKNN search, distance computation is the core task that dominates the runtime. Existing approaches typically use approximate distances to improve computational efficiency, often at the cost of reduced search accuracy. To address this issue, the state-of-the-art method, ADSampling, employs random projections to estimate approximate distances and introduces an additional distance correction process to mitigate accuracy loss. However, ADSampling has limitations in both effectiveness and generality, primarily due to its reliance on random projections for distance approximation and correction. To address the effectiveness limitations of ADSampling, we leverage data distribution to improve distance computation via orthogonal projection. Furthermore, to overcome the generality limitations of ADSampling, we adopt a data-driven approach to distance correction, decoupling the correction process from the distance approximation process. Extensive experiments demonstrate the superiority and effectiveness of our method. In particular, compared to ADSampling, our method achieves a speedup of 1.6 to 2.1 times on real-world datasets while providing higher accuracy.

Worst-case Performance of Popular Approximate Nearest Neighbor Search Implementations: Guarantees and Limitations

Abstract:Graph-based approaches to nearest neighbor search are popular and powerful tools for handling large datasets in practice, but they have limited theoretical guarantees. We study the worst-case performance of recent graph-based approximate nearest neighbor search algorithms, such as HNSW, NSG and DiskANN. For DiskANN, we show that its "slow preprocessing" version provably supports approximate nearest neighbor search query with constant approximation ratio and poly-logarithmic query time, on data sets with bounded "intrinsic" dimension. For the other data structure variants studied, including DiskANN with "fast preprocessing", HNSW and NSG, we present a family of instances on which the empirical query time required to achieve a "reasonable" accuracy is linear in instance size. For example, for DiskANN, we show that the query procedure can take at least $0.1 n$ steps on instances of size $n$ before it encounters any of the $5$ nearest neighbors of the query.

Abstract:The Closest Pair Problem (CPP) is one of the fundamental problems that has a wide range of applications in data mining, such as unsupervised data clustering, user pattern similarity search, etc. A number of exact and approximate algorithms have been proposed to solve it in the low dimensional space. In this paper, we address the problem when the metric space is of a high dimension. For example, the drug-target or movie-user interaction data could contain as many as hundreds of features. To solve this problem under the (ell _2) norm, we present two novel approximate algorithms. Our algorithms are based on the novel idea of projecting the points into the real line. We prove high probability bounds on the run time and accuracy for both of the proposed algorithms. Both algorithms are evaluated via comprehensive experiments and compared with existing best-known approaches. The experiments reveal that our proposed approaches outperform the existing methods.

Abstract:Locality sensitive hashing (LSH) and its variants are widely used for approximate kNN (k nearest neighbor) search in high-dimensional space. The success of these techniques largely depends on the ability of preserving kNN information. Unfortunately, LSH only provides a high probability that nearby points in the original space are projected into nearby region in a new space. This potentially makes many false positives and false negatives resulting from unrelated points. Many extensions of LSH aim to alleviate the above issue by improving the distance preserving ability. In this paper, we abound improving LSH function but propose a novel idea to enhance the performance by transforming the original data to a new space before applying LSH. A preserving-ignoring transformation (PIT) function satisfying some rigorous conditions can be used to convert original points to an interim space with strict distance preserving-ignoring capacity. Based on this property, a linear order is utilized to build an efficient index structure in the interim space. Finally, LSH can be applied to candidate set searched by our index structure for final results. Experiments are conducted and the proposed approach performs better than state-of-the-art methods SK-LSH, DSH and NSH in terms of both accuracy and efficiency.

Abstract:Nearest neighbor search is a fundamental and essential operation in applications from many domains, such as databases, machine learning, multimedia, and computer vision. Because exact searching results are not efficient for a high-dimensional space, a lot of efforts have turned to approximate nearest neighbor search. Although many algorithms have been continuously proposed in the literature each year, there is no comprehensive evaluation and analysis of their performance. In this paper, we conduct a comprehensive experimental evaluation of many state-of-the-art methods for approximate nearest neighbor search. Our study (1) is cross-disciplinary (i.e., including 19 algorithms in different domains, and from practitioners) and (2) has evaluated a diverse range of settings, including 20 datasets, several evaluation metrics, and different query workloads. The experimental results are carefully reported and analyzed to understand the performance results. Furthermore, we propose a new method that achieves both high query efficiency and high recall empirically on majority of the datasets under a wide range of settings.

Abstract:Nowadays, Nearest Neighbor Search becomes more and more important when facing the challenge of big data. Traditionally, to solve this problem, researchers mainly focus on building effective data structures such as hierarchical k -means tree or using hashing methods to accelerate the query process. In this paper, we propose a novel unified approximate nearest neighbor search scheme to combine the advantages of both the effective data structure and the fast Hamming distance computation in hashing methods. In this way, the searching procedure can be further accelerated. Computational complexity analysis and extensive experiments have demonstrated the effectiveness of our proposed scheme.

Abstract:Due to the "curse of dimensionality" problem, it is very expensive to process the nearest neighbor (NN) query in high dimensional spaces; and hence, approximate approaches, such as Locality-Sensitive Hashing (LSH), are widely used for their theoretical guarantees and empirical performance. Current LSH-based approaches target at the l(1) and l(2) spaces, while as shown in previous work, the fractional distance metrics (l(p) metrics with 0 < p < 1) can provide more insightful results than the usual l(1) and l(2) metrics for data mining and multimedia applications. However, none of the existing work can support multiple fractional distance metrics using one index. In this paper, we propose LazyLSH that answers approximate nearest neighbor queries for multiple l(p) metrics with theoretical guarantees. Different from previous LSH approaches which need to build one dedicated index for every query space, LazyLSH uses a single base index to support the computations in multiple l(p) spaces, significantly reducing the maintenance overhead. Extensive experiments show that LazyLSH provides more accurate results for approximate kNN search under fractional distance metrics.

Abstract:Recent years have witnessed growing interests in computing compact binary codes and binary visual descriptors to alleviate the heavy computational costs in large-scale visual research. However, it is still computationally expensive to linearly scan the large-scale databases for nearest neighbor NN search. In [15], a new approximate NN search algorithm is presented. With the concept of bridge vectors which correspond to the cluster centers in Product Quantization [10] and the augmented neighborhood graph, it is possible to adopt an extract-on-demand strategy on the online querying stage to search with priority. This paper generalizes the algorithm to the Hamming space with an alternative version of k-means clustering. Despite the simplicity, our approach achieves competitive performance compared to the state-of-the-art methods, i.e., MIH and FLANN, in the aspects of search precision, accessed data volume and average querying time.

Abstract:Locality sensitive hashing LSH is the most popular algorithm for approximate nearest neighbor ANN search. As LSH partitions vector space uniformly and the distribution of vectors is usually non-uniform, it poorly fits real dataset and has limited performance. In this paper, we propose a new data-dependent LSH algorithm, which has two-level structures to perform ANN search in high dimensional spaces. In the first level, we first train a number of cluster centers, then use the cluster centers to divide the dataset into many clusters and the vectors in each cluster has near uniform distribution. In the second level, we construct LSH tables for each cluster. Given a query, we first determine a few clusters that it belongs to with high probability, and then perform ANN search in the corresponding LSH tables. Experimental results on the reference datasets show that the search speed can be increased by 48 times compared to E2LSH, while keeping high search precision.
Discovering Data Structures: Nearest Neighbor Search and Beyond

Abstract:We propose a general framework for end-to-end learning of data structures. Our framework adapts to the underlying data distribution and provides fine-grained control over query and space complexity. Crucially, the data structure is learned from scratch, and does not require careful initialization or seeding with candidate data structures/algorithms. We first apply this framework to the problem of nearest neighbor search. In several settings, we are able to reverse-engineer the learned data structures and query algorithms. For 1D nearest neighbor search, the model discovers optimal distribution (in)dependent algorithms such as binary search and variants of interpolation search. In higher dimensions, the model learns solutions that resemble k-d trees in some regimes, while in others, they have elements of locality-sensitive hashing. The model can also learn useful representations of high-dimensional data and exploit them to design effective data structures. We also adapt our framework to the problem of estimating frequencies over a data stream, and believe it could also be a powerful discovery tool for new problems.

Abstract:We prove an $\Omega(d/\log \frac{sw}{nd})$ lower bound for the average-case cell-probe complexity of deterministic or Las Vegas randomized algorithms solving approximate near-neighbor (ANN) problem in $d$-dimensional Hamming space in the cell-probe model with $w$-bit cells, using a table of size $s$. This lower bound matches the highest known worst-case cell-probe lower bounds for any static data structure problems. This average-case cell-probe lower bound is proved in a general framework which relates the cell-probe complexity of ANN to isoperimetric inequalities in the underlying metric space. A tighter connection between ANN lower bounds and isoperimetric inequalities is established by a stronger richness lemma proved by cell-sampling techniques.

Abstract:We propose a novel approach to solving the approximate k-nearest neighbor search problem in metric spaces. The search structure is based on a navigable small world graph with vertices corresponding to the stored elements, edges to links between them, and a variation of greedy algorithm for searching. The navigable small world is created simply by keeping old Delaunay graph approximation links produced at the start of construction. The approach is very universal, defined in terms of arbitrary metric spaces and at the same time it is very simple. The algorithm handles insertions in the same way as queries: by finding approximate neighbors for the inserted element and connecting it to them. Both search and insertion can be done in parallel requiring only local information from the structure. The structure can be made distributed. The accuracy of the probabilistic k-nearest neighbor queries can be adjusted without rebuilding the structure.The performed simulation for data in the Euclidean spaces shows that the structure built using the proposed algorithm has small world navigation properties with log2(n) insertion and search complexity at fixed accuracy, and performs well at high dimensionality. Simulation on a CoPHiR dataset revealed its high efficiency in case of large datasets (more than an order of magnitude less metric computations at fixed recall) compared to permutation indexes. Only 0.03% of the 10 million 208-dimensional vector dataset is needed to be evaluated to achieve 0.999 recall (virtually exact search). For recall 0.93 processing speed 2800queries/s can be achieved on a dual Intel X5675 Xenon server node with Java implementation.

Abstract:Binary hashing has been widely studied for approximate nearest neighbor ANN search with its compact representation and efficient comparison. Many existing hashing methods aim at improving the accuracy of ANN search, but ignore the complexity of generating binary codes. In this paper, we propose a new unsupervised hashing method based on a sparse matrix, named as Sparse Matrix based Hashing SMH. There are only three kinds of elements in our sparse matrix, i.e., +1, $$-1$$-1 and 0. We learn the sparse matrix by optimizing a new pair-wise distance-preserving objective, in which the linear projection on the Euclidean distance and the corresponding Hamming distance is preserved. With the special form of the sparse matrix, the optimization can be solved by a greedy algorithm. The experiments on two large-scale datasets demonstrate that SMH expedites the process of generating binary codes, and achieves competitive performance with the state-of-the-art unsupervised hashing methods.
Efficient Data-aware Distance Comparison Operations for High-Dimensional Approximate Nearest Neighbor Search

Abstract:High-dimensional approximate $K$ nearest neighbor search (AKNN) is a fundamental task for various applications, including information retrieval. Most existing algorithms for AKNN can be decomposed into two main components, i.e., candidate generation and distance comparison operations (DCOs). While different methods have unique ways of generating candidates, they all share the same DCO process. In this study, we focus on accelerating the process of DCOs that dominates the time cost in most existing AKNN algorithms. To achieve this, we propose an \underline{D}ata-\underline{A}ware \underline{D}istance \underline{E}stimation approach, called \emph{DADE}, which approximates the \emph{exact} distance in a lower-dimensional space. We theoretically prove that the distance estimation in \emph{DADE} is \emph{unbiased} in terms of data distribution. Furthermore, we propose an optimized estimation based on the unbiased distance estimation formulation. In addition, we propose a hypothesis testing approach to adaptively determine the number of dimensions needed to estimate the \emph{exact} distance with sufficient confidence. We integrate \emph{DADE} into widely-used AKNN search algorithms, e.g., \emph{IVF} and \emph{HNSW}, and conduct extensive experiments to demonstrate the superiority.

Subspace Collision: An Efficient and Accurate Framework for High-dimensional Approximate Nearest Neighbor Search

Abstract:Approximate Nearest Neighbor (ANN) search in high-dimensional Euclidean spaces is a fundamental problem with a wide range of applications. However, there is currently no ANN method that performs well in both indexing and query answering performance, while providing rigorous theoretical guarantees for the quality of the answers. In this paper, we first design SC-score, a metric that we show follows the Pareto principle and can act as a proxy for the Euclidean distance between data <a class="link-external link-http" href="http://points.Inspired" rel="external noopener nofollow">this http URL</a> by this, we propose a novel ANN search framework called Subspace Collision (SC), which can provide theoretical guarantees on the quality of its results. We further propose SuCo, which achieves efficient and accurate ANN search by designing a clustering-based lightweight index and query strategies for our proposed subspace collision framework. Extensive experiments on real-world datasets demonstrate that both the indexing and query answering performance of SuCo outperform state-of-the-art ANN methods that can provide theoretical guarantees, performing 1-2 orders of magnitude faster query answering with only up to one-tenth of the index memory footprint. Moreover, SuCo achieves top performance (best for hard datasets) even when compared to methods that do not provide theoretical guarantees. This paper was published in SIGMOD 2025.
