Abstract:This paper addresses the problem of a single rumor source detection with multiple observations, from a statistical point of view of a spreading over a network, based on the susceptible-infectious model. For tree networks, multiple sequential observations for one single instance of rumor spreading cannot improve over the initial snapshot observation. The situation dramatically improves for multiple independent observations. We propose a unified inference framework based on the union rumor centrality, and provide explicit detection performance for degree-regular tree networks. Surprisingly, even with merely two observations, the detection probability at least doubles that of a single observation, and further approaches one, i.e., reliable detection, with increasing degree. This indicates that a richer diversity enhances detectability. For general graphs, a detection algorithm using a breadth-first search strategy is also proposed and evaluated. Besides rumor source detection, our results can be used in network forensics to combat recurring epidemic-like information spreading such as online anomaly and fraudulent email spams.

Abstract:This paper studies the problem of a single rumor source detection based on the susceptible-infected-susceptible (SIS) spreading model. Based on the rumor centrality proposed in the Susceptible-Infected (SI) model by Shah and Zaman, we propose a rumor centrality based algorithm, that leverages multiple observations to first construct a diffusion tree graph, and then use the union rumor centrality to find the rumor source. Our simulation results on different network structures shows that our proposed algorithm performs well. For tree networks, increasing the observations can dramatically improve the exact detection probability. This clearly indicates that a richer diversity enhances detect-ability.

Abstract:Identifying sources of epidemic spreading or rumor diffusion from minority data is of paramount importance in network science with great applied values to the society. However, a general theoretical frame work dealing with source(s) localization is lacking of perfect understanding. Based on limited observers in the network, we study the problem of estimating the origin of a disease/rumor outbreak: given a contact network and a snapshot of epidemic spread at a certain time, root out the infection source. Assuming that the epidemic spread follows the usual susceptible-infected (SI) model, we introduce an inference algorithm based on sparsely placed observers. We present an algorithm which utilizes the correlated information between the network structure (shortest paths) and the diffusion dynamics (time sequence of infection). The numerical results of artificial and empirical networks show that it leads to significant improvement of performance compared to existing approaches. Our analysis sheds insight into the behavior of the disease/rumor spreading process not only in the local particular regime but also for the whole general network. (C) 2019 Elsevier B.V. Abstract:The openness characteristic of social networks facilitates the rapid spread of rumors, necessitating effective methods for detecting and managing the abundance of rumors on social media. Existing studies have primarily focused on improving the accuracy of rumor detection, but often overlook the vital aspects of interpretability and explanation of rumor patterns, limiting their credibility and real-world usability. Additionally, previous works have typically examined only a subset of user features, content, and spreading structure, neglecting the analysis of compound rules. To address these limitations, we propose a novel framework for detecting rumor patterns that emphasize comprehensive feature construction and the explanation of compound rules. Our framework incorporates multi-dimensional features, including user characteristics, post content, and the structure of information propagation. Advanced techniques, including large language models (such as ChatGPT) and graph motif discovery algorithms, are employed for feature construction. By leveraging diverse features, crucial integrated rules identified by Rulefit can investigate the contextually dependent associations among various interrelated rumor factors. We consolidate and analyze seven distinct rumor patterns based on the Credible Early Detection Dataset, deriving valuable insights into the inherent characteristics of rumors. The recognition of rumor patterns empowers social media platforms and fact-checking organizations to develop targeted and explainable interventions that effectively mitigate the spread of rumors and safeguard the integrity of information. These interventions greatly enhance the transparency and trustworthiness of rumor management, fostering a more reliable information ecosystem.

Abstract:Suppose that a rumor originating from a single source among a set of suspects spreads in a network, how to root out this rumor source? With the a priori knowledge of suspect nodes and an observation of infected nodes, we construct a maximum a posteriori (MAP) estimator to identify the rumor source using the susceptible-infected (SI) model. The a priori suspect set and its associated connectivity bring about new ingredients to the problem, and thus we propose to use local rumor center, a generalized concept based on rumor centrality, to identify the source from suspects. For regular tree-type networks of node degree {\delta}, we characterize Pc(n), the correct detection probability of the estimator upon observing n infected nodes, in both the finite and asymptotic regimes. First, when every infected node is a suspect, Pc(n) asymptotically grows from 0.25 to 0.307 with {\delta} from 3 to infinity, a result first established in Shah and Zaman (2011, 2012) via a different approach; and it monotonically decreases with n and increases with {\delta}. Second, when the suspects form a connected subgraph of the network, Pc(n) asymptotically significantly exceeds the a priori probability if {\delta}>2, and reliable detection is achieved as {\delta} becomes large; furthermore, it monotonically decreases with n and increases with {\delta}. Third, when there are only two suspects, Pc(n) is asymptotically at least 0.75 if {\delta}>2; and it increases with the distance between the two suspects. Fourth, when there are multiple suspects, among all possible connection patterns, that they form a connected subgraph of the network achieves the smallest detection probability. Our analysis leverages ideas from the Polya's urn model in probability theory and sheds insight into the behavior of the rumor spreading process not only in the asymptotic regime but also for the general finite-n regime.

Abstract:Identifying rumor sources in online social networks (OSNs) plays a crucial role in controlling the spread of rumors and mitigating their damage. However, the community structure of OSNs and timeliness of rumors increase the complexity of accurately characterizing rumor-spreading behavior, making it extremely challenging to identify the source of rumor in OSNs. Conventional studies on rumor source identification often overlook the community structure of OSNs and timeliness of rumors. This paper proposes a rumor sources identification framework that take these two aspects into consideration. First, we transfer the snapshots of a dynamic OSN into a community-structured dynamic OSN through 4 meticulously designed phases. Second, instead of considering a constant influence of rumors in traditional techniques, we introduce a time-varying dynamic propagation parameter to quantify the timeliness of rumor, and apply the propagation parameter to establish a microscopic rumor spreading model. This process addresses the issue of modeling the timeliness of rumor. Third, we adopt sensor-based observation techniques to collect the propagation information of rumor, and a hybrid sensor deployment strategy is designed to improve the efficiency of information collection. Fourth, we propose an algorithm for identifying single and multiple rumor sources in community-structured dynamic OSN, this algorithm initiates with the utilization of some criteria to analyze the gathered propagation information and estimate the suspicious communities that harbor the source of rumors. Subsequently, it applies maximum likelihood estimation method within each community to determine the ultimate source of the rumor. Experimental results on real-world and synthetic networks indicate that our method can accurately identify the real rumor sources. To the best of our knowledge, the proposed method is the first that can be used to identify rumor sources in community-structured dynamic OSNs.

Abstract:Rumor spreading has been studied for decades, but its underlying mechanism is still under debate, especially for those ones based on internet. By focusing on the spreading data of six typical events on Sina Weibo, we surprisingly find that the spreading of modern news shows some new features, i.e. either explosively fast or slow, depending on the individual events. To understand its mechanism, we present a Susceptible-Accepted-Recovered (SAR) model with both information sensitivity and social reinforcement. By numerical simulations we show that the model can reproduce the main spreading patterns of the six typical events and the spreading speed can be promoted by increasing either the strength of information sensitivity or the social reinforcement. Moreover, we find that the dependence of final accepted size on some key parameters, such as the transmission probability and information sensitivity, can change from continuous to discontinuous when the strength of the social reinforcement is large. An edge-based theory analysis is presented to explain the explosive spreading by information sensitivity and social reinforcement.

Abstract:We consider the problem of identifying rumor sources in a network, in which rumor spreading obeys a time-slotted susceptible-infected model. Unlike existing approaches, our proposed algorithm identifies as sources those nodes, which when set as sources, result in the smallest dominant eigenvalue of the corresponding reduced nonbacktracking matrix deduced from message passing equations. We also propose a reduced-complexity algorithm derived from the previous algorithm through a perturbation approximation. Numerical experiments on synthesized and real-world networks suggest that these proposed algorithms generally have higher accuracy compared with representative existing algorithms.

Abstract:We provide a systematic study of the problem of finding the source of a rumor in a network. We model rumor spreading in a network with the popular susceptible-infected (SI) model and then construct an estimator for the rumor source. This estimator is based upon a novel topological quantity which we term rumor centrality. We establish that this is a maximum likelihood (ML) estimator for a class of graphs. We find the following surprising threshold phenomenon: on trees which grow faster than a line, the estimator always has nontrivial detection probability, whereas on trees that grow like a line, the detection probability will go to 0 as the network grows. Simulations performed on synthetic networks such as the popular small-world and scale-free networks, and on real networks such as an internet AS network and the U.S. electric power grid network, show that the estimator either finds the source exactly or within a few hops of the true source across different network topologies. We compare rumor centrality to another common network centrality notion known as distance centrality. We prove that on trees, the rumor center and distance center are equivalent, but on general networks, they may differ. Indeed, simulations show that rumor centrality outperforms distance centrality in finding rumor sources in networks which are not tree-like.

Information Source Detection Via Maximum A Posteriori Estimation

Abstract:The problem of information source detection, whose goal is to identify the source of a piece of information from a diffusion process (e.g., computer virus, rumor, epidemic, and so on), has attracted ever-increasing attention from research community in recent years. Although various methods have been proposed, such as those based on centrality, spectral and belief propagation, the existing solutions still suffer from high time complexity and inadequate effectiveness. To this end, we revisit this problem in the paper and present a comprehensive study from the perspective of likelihood approximation. Different from many previous works, we consider both infected and uninfected nodes to estimate the likelihood for the detection. Specifically, we propose a Maximum A Posteriori (MAP) estimator to detect the information source for general graphs with rumor centrality as the prior. To further improve the efficiency, we design two approximate estimators, namely Brute Force Search Approximation (BFSA) and Greedy Search Bound Approximation (GSBA). BFSA tries to traverse the permitted permutations and directly computes the likelihood, while GSBA exploits a strategy of greedy search to find a surrogate upper bound of the probabilities of permitted permutations for a given node, and derives an approximate MAP estimator. Extensive experiments on several network data sets clearly demonstrate the effectiveness of our methods in detecting the single information source.
Early Detection of Rumors in Heterogeneous Mobile Social Network.

Abstract:Online rumors may stimulate the diffusion of misinformation in the social network or even panic among people. The rapid development of mobile social network (MSN) provides a favourable environment for the rumors to be widely spread. Previous research mainly focuses on detecting the rumor in the interest-based social network and designing mechanisms to minimize the diffusion of rumors. However, many proposals for interest-based social network will not work well in MSN, due to the fact that few lexicon features can be extracted through MSN. In this paper, we analyze the structure of the information diffusion graph of MSN, and propose a diffusion model to explain the spread of information in MSN. As the MSN can be treated as a heterogeneous network, we design an algorithm to learn the latent factors of each piece of information. The learned factors can be leveraged to detect the rumors. Experiments on a real-world MSN dataset show that our proposed algorithm outperforms other approaches, and can reach 61% on the precision metric.
Precise Modeling Rumor Propagation and Control Strategy on Social Networks

Abstract:In this paper, we first point out the limitations of the classic epidemic spreading model SIR in representing rumor spreading processes, and then identify the effect of public opinions in dividing Infected states (I) into Positive infected (P) states and Negative infected (N) states. Based on this observation, we propose a new SPNR model. To evaluate the proposed model, we compare the simulation results with the real-world data obtained on Sina Weibo, the largest micro-blogging tool in China. The results show that the new model effectively captures the rumor spreading process. Furthermore, to develop an effective rumor control strategy, we propose an opinion guidance rumor control strategy based on SPNR model. We compare different control strategies using real-world data sets and a synthetic network generated according to a scale-free model. The results show that the proposed strategy is effective in fighting rumor spreading.

Abstract:With the increasing popularity of mobile devices, each user is able to conveniently acquire messages from others, and share diverse forms of information, like texts, images, or videos through online mobile apps. The full freedom of speech makes a great amount of truth (i.e., true information) and rumor (i.e., false information) propagate rapidly in a hybrid way through mobile platforms. As a huge variety of information floods pouring over us each day, identifying the authenticity of massive events becomes a necessary task to maintain the stability of Mobile Social Networks (MSNs). An important way to realize it is to trace their diffusions and make judgements according to the reliability of sources. With this regard, this paper proposes a diffusion model that characterizes the simultaneous diffusion of both truth and rumor in realistic MSNs, and makes the first attempt to figure out their respective sources. The problem of interest can be stated as: Given an outcome of cascade of both truth and rumor in MSNs, i.e., a set of nodes that might be the ignorant, the spreader of truth or rumor, or simply the silent receiver, how can we infer both truth sources and rumor sources? Different from previous sources detection works considering single type of nodes, the interplay between truth diffusions and rumor diffusions makes the conventional methods not work. To answer this question, we aim to maximize the similarity index, i.e., the number of nodes possessing the same states between the resulting network triggered by our estimated sources with the proposed diffusion model and the given observation network. Compared with existing techniques to trace diffusions of truth or rumor, it is much harder to find two kinds of sets at the same time, including truth sources and rumor sources, due to two primary reasons: (i) our biset optimization makes the submodularity techniques fail; (ii) our objective function is proven to be non-bisubmodular. To overcome above limitations, we first convert the objective similarity index into a bisubmodular function by virtue of set covering. Based on this, we propose an approximation algorithm called Truth and Rumor Sources Detection (TRSD) algorithm via multiple reverse samplings with a provable $\frac{1}{4(1+\epsilon)^2}$14(1+ε)2 approximation ratio. Further, a novel “time reversal” sources optimization strategy is proposed to converge the number of output sources from TRSD to a steady state. The effectiveness of our models and algorithms are empirical validated in two various datasets, from which we observe an up to 15% of similarity index gain as well as a narrowed down gap 0.6% to the ground truth.

Abstract:The history of rumors might be as long as the history of human beings. Not much is known about this phenomenon until very recently when social networks provide a more efficient way for online rumor spreading. Microblogging platform, like Twitter and Sina Weibo, provides an ideal environment not only for rumor spreading, but also fruitful data to reveal the underlying rules controlling the birth, spread, and death of rumors. In this paper, we try to answer the following questions which have been confusing people for years. How do rumor propagate in the network? How do human factors affect the spreading patterns of rumor? How do we construct models to understand the collective group behavior based on probabilistic individual choices? Our study on microblogging systems help to expose the digital traces of online rumor spreading, which offers an opportunity to investigate how netizens interact with each other in the process of rumor spreading. Based on the analysis of the interactions, we propose a mathematical model running on real topologies to simulate this process and explore the characteristics of online rumor spreading. Experiments show that our model can reflect the transmission pattern of real rumors. Our work is different from previous ones by pointing out that a subset of the population can work as "Resisters" who are proactively persuading their neighbors not to believe the rumor, while previous works only label them as the "silent" nodes. To the best of our knowledge, this is the first time to emphasize the contribution of "Resisters" and to mathematically study their influence on the rumor spreading process.

Abstract:Rumor diffusion on complex networks has been widely investigated assuming that an individual learns the rumor merely from its neighbors, which, however, is not always the case. Recent studies of layered models have shown that individuals belonging to many different networks can affect the spreading process on one network. In this paper, we take this phenomenon into consideration and discuss its influence on rumor diffusion in complex networks by introducing independent spreaders. Independent spreaders are nodes that know the rumor from other channels rather than their neighbors. A new stochastic technique is used to obtain the dynamics of rumor diffusion. Results reveal that independent spreaders boost the process by bringing the rumor to regions remote from current spreaders. In order to accelerate diffusion, we find that improving the network connectivity is more efficient than adding more independent spreaders.

Abstract:Social media platforms are broadly used to exchange information by milliards of people worldwide. Each day people share a lot of their updates and opinions on various types of topics. Moreover, politicians also use it to share their postulates and programs, shops to advertise their products, etc. Social media are so popular nowadays because of critical factors, including quick and accessible Internet communication, always available. These conditions make it easy to spread information from one user to another in close neighborhoods and around the whole social network located on the given platform. Unfortunately, it has recently been increasingly used for malicious purposes, e.g., rumor propagation. In most cases, the process starts from multiple nodes (users). There are numerous papers about detecting the real source with only one initiator. There is a lack of solutions dedicated to problems with multiple sources. Most solutions that meet those criteria need an accurate number of origins to detect them correctly, which is impossible to obtain in real-life usage. This paper analyzes the methods to detect rumor outbreaks in online social networks that can be used as an initial guess for the number of real propagation initiators.
