This big data can be useful in identifying safety hazardous zones, which can be complicated and unreliable today. Without sufficient data, past studies had to focus mostly on the micro level networks. Research on macro-level hotzone identification is limited, and until this point, the contribution of various macroscopic features on the macro-level crash risks is still in dispute. This paper, with the help of massive amount of data, investigates the feasibility of using random forest for hotzone identification at macro-level- the Traffic Analysis Zone (TAZ) level. At the same time, the most influential macro-level crash risk determinants were identified by applying a series of random forest models in combination with the cross validation methods. The differences of all features between hotzones and normal TAZs were also recognized through Wilcoxon tests. Crash data of three counties in Florida during 2008 and 2009 were employed. Crash risks by different injury levels and collision types were investigated separately. Finally, the significance of various macroscopic variables was determined by different types of crash risks using variable importance analysis.The research results suggest that the distribution of road network and socio-economics are the two most important factors when proactively alleviating traffic safety issues. For developed urban areas, it is desirable to formulate specific traffic safety management strategies that accounts for zone-level socioeconomics and development of road infrastructure. For zones with a higher percentage of school enrollment, pedestrian and bicycle friendly roadway system design are most beneficial. It is also desirable to take efficient countermeasures such as law enforcement and driving school training to regulate young drivers' behavior in school zones. For areas with high minority residence, there might be a need to use awareness campaigns in multiple languages to relieve pedestrian safety issues. Finally, additional attention should be paid to improve intersection design and management during the planning and operation processes. Published by Elsevier B.V.
Characteristic of macroscopic fundamental diagrams based on mobile sensing data

Abstract:An approach to reconstruct the macroscopic fundamental diagram (MFD) was proposed based on probe data in order to detect and evaluate the congestion of urban traffic network in real time ,and analyze the inherent characteristic of urban traffic flow on road network .The characteristics and variation patterns of MFD were analyzed .Given the non-homogeneous distribution of probe penetration rates ,procedures were presented to magnify MFD variables with varying penetration rates estimated by the GPS data combined with the fixed detections .The accuracy and the characteristic of MFD were tested with trajectories of 7 109 taxis in Hangzhou , China.An estimation method of expansion coefficients was presented for the MFD reconstruction ,using piecewise mean according to the ranges of the flow rate and density ,respectively .The method generates a more accurate MFD that can be useful to inform real-time traffic monitoring required to implement control strategies in the field compared with the historical mean as the uniform expansion coefficient .
Cellular Signaling Data Driven Simulation-Based Dynamic Traffic Assignment and Its Applications to a Real-World Road Network

Abstract:This paper presents a big data driven simulation-based dynamic traffic assignment (DTA) model by combining cellular signaling data, remote microwave sensors and license plate recognition (LPR) cameras data. First, the static origin destination (OD) matrix is estimated by using cellular signaling data. Second, remote microwave and LPR data are fused to calibrate parameters on the network supply side, including the link fundamental diagram calibration and link impedance function calibration. Third, a mesoscopic simulation model is developed by using DTALite, and the dynamic OD calibration is conducted by comparing link flows generated by simulation-based DTA and measured by remote microwave sensors. Finally, this paper takes the real-world road network of Hangzhou as an example to quantitatively assess impacts of large-scale implemented work zones before the 2016 G20 Summit and adverse weather conditions on the road network performance with the developed model. Results show the big data driven simulation-based DTA model developed in this paper has wide prospects of applications in the evaluation and optimization of comprehensive transportation management strategies.
Hotspot identification considering daily variability of traffic flow and crash record: A case study

Abstract:Hotspots identification (HSID), a reactive crash prediction based on the historical accident counts, is crucial to transport authorities for evaluating the risk level of the object road sites. The objective of the research is to identify unidentified hotspots that should have been treated. Numerous conventional HSID approaches have been developed and applied for decades, none of which takes daily variability of traffic flow and crash record into account. In this regard, we categorize the time of day into four groups: (1) morning peak hours, (2) afternoon peak hours, (3) daytime, and (4) night off-peak hours. The authors further apply this proposed methodology to Pacific Motorway Southeast Queensland section linking Brisbane to Gold Coast based on an Empirical Bayesian (EB) approach. Finally, the applications of these proposed EB-based methods and the conventional EB method are discussed through an aggregated view.

Abstract:Zonal crash prediction has been one of the most prevalent topics in recent traffic safety research. Typically, zonal safety level is evaluated by relating aggregated crash statistics at a certain spatial scale to various macroscopic factors. Another potential solution is from the micro level perspective, in which zonal crash frequency is estimated by summing up the expected crashes of all the road entities located within the zones of interest. This study intended to compare these two types of zonal crash prediction models. The macro-level Bayesian spatial model with conditional autoregressive prior and the micro-level Bayesian spatial joint model were developed and empirically evaluated, respectively. An integrated hot zone identification approach was then proposed to exploit the merits of separate macro and micro screening results. The research was based on a three-year dataset of an urban road network in Hillsborough County, Florida, U.S.Results revealed that the micro-level model has better overall fit and predictive performance, provides better insights about the micro factors that closely contribute to crash occurrence, and leads to more direct countermeasures. Whereas the macro-level crash analysis has the advantage of requirement of less detailed data, providing additional instructions for non-traffic engineering issues, as well as serving as an indispensable tool in incorporating safety considerations into long term transportation planning. Based on the proposed integrated screening approach, specific treatment strategies could be proposed to different screening categories. Leveraging Connected Vehicle Data for Near-Crash Detection and Analysis in Urban Environments

Abstract:Urban traffic safety is a pressing concern in modern transportation systems, especially in rapidly growing metropolitan areas where increased traffic congestion, complex road networks, and diverse driving behaviors exacerbate the risk of traffic incidents. Traditional traffic crash data analysis offers valuable insights but often overlooks a broader range of road safety risks. Near-crash events, which occur more frequently and signal potential collisions, provide a more comprehensive perspective on traffic safety. However, city-scale analysis of near-crash events remains limited due to the significant challenges in large-scale real-world data collection, processing, and analysis. This study utilizes one month of connected vehicle data, comprising billions of records, to detect and analyze near-crash events across the road network in the City of San Antonio, Texas. We propose an efficient framework integrating spatial-temporal buffering and heading algorithms to accurately identify and map near-crash events. A binary logistic regression model is employed to assess the influence of road geometry, traffic volume, and vehicle types on near-crash risks. Additionally, we examine spatial and temporal patterns, including variations by time of day, day of the week, and road category. The findings of this study show that the vehicles on more than half of road segments will be involved in at least one near-crash event. In addition, more than 50% near-crash events involved vehicles traveling at speeds over 57.98 mph, and many occurred at short distances between vehicles. The analysis also found that wider roadbeds and multiple lanes reduced near-crash risks, while single-unit trucks slightly increased the likelihood of near-crash events. Finally, the spatial-temporal analysis revealed that near-crash risks were most prominent during weekday peak hours, especially in downtown areas.

Abstract:VANETs enable information exchange among vehicles, other end devices and public networks, which plays a key role in road safety/infotainment, intelligent transportation systems, and self-driving systems. As vehicular connectivity soars, and new on-road mobile applications and technologies emerge, VANETs are generating an ever-increasing amount of data, requiring fast and reliable transmissions through VANETs. On the other hand, a variety of VANETs related data can be analyzed and utilized to improve the performance of VANETs. In this article, we first review VANETs technologies to efficiently and reliably transmit big data. Then, the methods employing big data for studying VANETs characteristics and improving VANETs performance are discussed. Furthermore, we present a case study where machine learning schemes are applied to analyze VANETs measurement data for efficiently detecting negative communication conditions.

Air Pollution Hotspot Detection and Source Feature Analysis using Cross-domain Urban Data

Abstract:Air pollution is a major global environmental health threat, in particular for people who live or work near pollution sources. Areas adjacent to pollution sources often have high ambient pollution concentrations, and those areas are commonly referred to as air pollution hotspots. Detecting and characterizing pollution hotspots are of great importance for air quality management, but are challenging due to the high spatial and temporal variability of air pollutants. In this work, we explore the use of mobile sensing data (i.e., air quality sensors installed on vehicles) to detect pollution hotspots. One major challenge with mobile sensing data is uneven sampling, i.e., data collection can vary by both space and time. To address this challenge, we propose a two-step approach to detect hotspots from mobile sensing data, which includes local spike detection and sample-weighted clustering. Essentially, this approach tackles the uneven sampling issue by weighting samples based on their spatial frequency and temporal hit rate, so as to identify robust and persistent hotspots. To contextualize the hotspots and discover potential pollution source characteristics, we explore a variety of cross-domain urban data and extract features from them. As a soft-validation of the extracted features, we build hotspot inference models for cities with and without mobile sensing data. Evaluation results using real-world mobile sensing air quality data as well as cross-domain urban data demonstrate the effectiveness of our approach in detecting and inferring pollution hotspots. Furthermore, the empirical analysis of hotspots and source features yields useful insights regarding neighborhood pollution sources.

Abstract:The development of social information technology provides technical support for the arrival of the big data era. Big data and its related technologies have been gradually integrated into people's lives. Conducting big data technology and data mining technology, this paper adopts the vehicle networking scheme in vehicle driving, that is, each vehicle is connected to a data center, and analyzes the driving safety on the basis of a large number of vehicle driving data. The algorithm can be subdivided into three steps: data acquisition, using time series analysis method to obtain driving indicators, and classification and processing of various indicators by clustering algorithm. Through data mining technology and driving safety algorithm, the risk factors in the process of vehicle driving can be found in time, so as to ensure vehicle driving safety.
A Spatial Autocorrelation-based Approach for Identifying Hot Spots on Urban Road

Abstract:An approach based on spatial autocorrelation analysis was presented to identify hot spots on urban road.The application of this methodology was illustrated by five-year's traffic crash data.Firstly,a non-parametric kernel density estimate sketched a model of two dimensional planar accident point spatial distribution.An estimation of the optimal bandwidth for accident distribution density was 115.2 m and subsequently was selected to create a spatial statistical unit on road segment.Then,the spatial statistical units were derived from a GIS-based region-arc topology model as a representation of the urban road network,and the attribute values of crash counts and severity indices were aggregated.Finally,the Globe Moran index was employed to examine spatial distribution clustered pattern of crash data.The local G-statistic was used to identify the clustering of low and high index values and to generate a crash hot spots map.Results of the research indicate that compared with the negative binomial model in modeling the crash frequency,the spatial analysis under integration of accident attribute data with position can not only identify hot spots on road segments(intersections) but also rank hot spots with spatial correlation according to the attribute values.Traffic management department can use the spatial analysis visualized results to locate hot spots and develop further traffic safety decision-making research.

Abstract:Road traffic crashes are common occurrences that create substantial losses and hazards to society. A complex interaction of components, including drivers, vehicles, roads, and the environment, can impact the causes of these crashes. Due to its complexity, crash identification, and prediction research over large-scale areas faces several obstacles, including high costs and challenging data collecting. This study offers a method for large-scale road network crash risk identification based on open-source data, given that roadways' horizontal and vertical geometric alignment is crucial in highway traffic crashes. This methodology includes a comprehensive technique for feature extraction from horizontal curves (H-curves) and vertical curves (V-curves) and a novel way of combining the XGBoost model's attributes with the Harris Hawks Optimization (HHO) algorithm-referred to as the HHO-XGBoost model. Using this model on the road geometry-crash risk dataset developed specifically for this study, the HHO approach adaptively identifies the optimal set of XGBoost hyperparameters and yields favorable outcomes. This study creates a three-dimensional road geometry database that may be utilized for various road infrastructure management, operation, and safety in addition to completing a tiered risk analysis of "region-road-segment" for large-scale road networks. It also offers direction on using swarm intelligence algorithms in integrated learning models.
Meso-level hotspot identification for suburban arterials.

Abstract:Accurate identification of crash hotspots forms the foundation of roadway safety improvement. The Highway Safety Manual micro-level approach uses individual intersections and road segments as analysis units, and correspondingly identifies some isolated road entities as hotspots. However, because traffic police and administrative agencies routinely conduct safety improvement based on multiple continuous segments and intersections, the identification of hotspots at the micro-level is inefficient for field application. To better meet this need, this study proposes a new meso-level approach to identify hotspots, specifically on suburban arterials. Meso-level analysis units of three different configurations (201, 150, and 100 units) were obtained by combining a set number of intersections and their adjacent segments according to crash distribution and homogeneity. Their influence areas were determined according to the proportion of urbanized land in areas perpendicularly adjacent to the arterials. Three Bayesian Poisson-lognormal conditional autoregressive models (PLN-CAR) considering spatial correlations were developed for each unit configuration, using the full Bayesian (FB) method to ameliorate random fluctuation in crash counts. Potential for safety improvement (PSI) values were calculated based on the modeling results and were used to identify hotspots. Two measures, i.e., the concentrated degree of hotspots (CDH) and the hotspot identification accuracy (HIA), were proposed to make a quantitative and comparative evaluation. Results showed that 1) arterials with more parallel roads suffer lower crash risk, and 2) considering both the hotspot distribution and the identification accuracy, the 150 meso-level unit configuration was the best. The proposed meso-level hotspot identification method promises to be adaptive to safety improvement practices on suburban arterials.
Network space analysis–based identification of road traffic accident hotspots: a case study

Abstract:This study proposed a method for identifying traffic accident (TA) hotspots. The method combines kernel density estimation (KDE) with network kernel density estimation (NKDE). The hotspots identified through NKDE can be overlaid on the high-risk areas (hot zones) identified using planar KDE, resulting in accurate hotspot identification. The research site was Zhenjiang City in Jiangsu Province, China; data on 410 fatal traffic accidents from 2017 to 2020 were collected. An average nearest neighbour (ANN) ratio (0.563) was obtained using the global auto nearest neighbour distance method; thus, the fatal TAs had a cluster-type distribution in the city. Subsequently, the maximum clustering distance (7812.842591 m) in the research site was analysed using Ripley's K-function, which yielded a reasonable KDE bandwidth and enabled identifying the distribution of hot zones for fatal TAs. Precise hotspot identification was achieved by overlaying the results of NKDE-based analysis in these hot zones. The proposed method was verified using data on 131 fatal TAs during January to July 2021. The results revealed that, in Zhenjiang City, the identification rate for hot zones and hotspots in hot zones was 71.75% and 38.29%, respectively, and the overall hotspot identification rate was 27.48%, demonstrating the method's ability to relatively accurately identify hotspot locations, information that can help traffic authorities implement preventive measures.

Analysis of Traffic Crashes Involving Pedestrians Using Big Data: Investigation of Contributing Factors and Identification of Hotspots

Abstract:This study aims to explore the potential of using big data in advancing the pedestrian risk analysis including the investigation of contributing factors and the hotspot identification. Massive amounts of data of Manhattan from a variety of sources were collected, integrated, and processed, including taxi trips, subway turnstile counts, traffic volumes, road network, land use, sociodemographic, and social media data. The whole study area was uniformly split into grid cells as the basic geographical units of analysis. The cell-structured framework makes it easy to incorporate rich and diversified data into risk analysis. The cost of each crash, weighted by injury severity, was assigned to the cells based on the relative distance to the crash site using a kernel density function. A tobit model was developed to relate grid-cell-specific contributing factors to crash costs that are left-censored at zero. The potential for safety improvement (PSI) that could be obtained by using the actual crash cost minus the cost of "similar" sites estimated by the tobit model was used as a measure to identify and rank pedestrian crash hotspots. The proposed hotspot identification method takes into account two important factors that are generally ignored, i.e., injury severity and effects of exposure indicators. Big data, on the one hand, enable more precise estimation of the effects of risk factors by providing richer data for modeling, and on the other hand, enable large-scale hotspot identification with higher resolution than conventional methods based on census tracts or traffic analysis zones.

Abstract:Abstract Inter-city highway plays an important role in modern urban life and generates sensory data with spatio-temporal characteristics. Its current situation and future trends are valuable for vehicles guidance and transportation security management. As a domain routine analysis, daily detection of traffic hotspots faces challenges in efficiency and precision, because huge data deteriorates processing latency and many correlative factors cannot be fully considered. In this paper, an ensemble-learning based method for potential traffic hotspots detection is proposed. Considering time, space, meteorology, and calendar conditions, daily traffic volume is modeled on heterogeneous data, and trends predictive error can be reduced through gradient boosting regression technology. Using real-world data from one Chinese provincial highway, extensive experiments and case studies show our methods with second-level executive latency with a distinct improvement in predictive precision.
How to Select the Appropriate Safety Measurement to Identify a Hotspot

Abstract:As the first and crucial step in improving the overall safety of a road network, hot spots identification (HSID) has been the focus of many research efforts. In general, most of the HSID methods employ either crash counts or crash rates to screen hazardous locations. However, there is a lack of empirical comparison of the two crash statistics in terms of their identification performances when dealing with HSID. To quantify the performance difference of the two crash statistics, both real road section accident data and experimentally derived simulated data are used in this paper. Three different tests are employed to evaluate different aspects of identification performance. Additionally, various levels of confidence are also explored across different situations. The results illustrate that crash counts significantly outperforms crash rates in identifying hot spots. The findings are in agreement with the other theoretical derivations shown in previous studies.

Abstract:Thermal imaging, when coupled with deep-learning-based analysis, can significantly improve highway work zone management and safety, though data scarcity in this field has been a historical challenge. We collected over 440 hours of thermal footage from highway sites in Massachusetts and New Hampshire and created a vehicle segmentation dataset featuring over 14,000 vehicle instances. We implement effective training strategies for deep learning models and develop algorithms to analyze vehicle trajectories and merging behaviors. Various visualization techniques are illustrated to better understand the extensive analytics data generated for each site, which can lead to development of data-driven strategies to improve traffic management and safety. Macro Level Safety Modeling and Impact Factor Analysis

Abstract:Due to the lack of systematic research for traffic safety at the planning stage,the relationship between macro level impact factors such as road network patterns,traffic features and other variables with transportation safety remains unclear,which leads to the shortage of available methods and tools to evaluate the safety of various transportation plans.Based on the data from the Orange County,Florida,this paper describes the system research on macro transportation safety modeling at traffic analysis zone(TAZ) level,Abstracting effective indices of road network patterns,traffic features and other macro level impact factors.Bayes Space Static Model was adopted to investigate the association between transportation safety and impact factors.Adjacent TAZs are always similar in economic development,road network structures,and traffic features;while TAZs located separately tend to be more diversity.Bayesian Conditional Autoregressive Regression(CAR) Models were used to analyze these spatial correlated data.Considering the different crash mechanisms of major roads and minor roads,new modeling strategy was proposed by modeling crashes on arterials and on local roads separately.The paper finds out there is a significant relationship between the road network patterns and safety,and the new modeling strategy is able to differentiate the safety effect for different types of crashes.
Hotspot identification on urban arterials at the meso level

Abstract:Urban arterials form the main structure of city street networks, and typically have high traffic volume and high crash frequency. To reduce the number of crashes, hotspot identification (HSID) is the first step in the traffic safety management process, and often utilizes crash prediction models. Classical crash prediction models investigate the relationship between roadway characteristics and traffic safety at the micro level, that is, they treat road segments and intersections as isolated units. Micro-level analysis has limitations, however, when examining urban arterial crashes: 1) signal spacing is typically short for urban arterials in dense street networks, and there are interactions between intersections and road segments that classical models do not accommodate; and 2) for practical engineering, a hotspot to which countermeasures are applied generally consists of several adjacent intersections and road segments instead of a single intersection or road segment. To address these concerns, signalized intersections and their adjacent road segments were combined into meso-level units, which were adopted to investigate traffic safety data from 21 urban arterials in Shanghai, China. To determine if the meso-level unit is the most suitable research unit for identifying hotspots on urban arterials, and if so, which HSID method can most consistently identify them, this study identified micro-level (separate intersection and road segment) and meso-level (combined intersection and road segment) hotspots using crash frequency, empirical Bayesian (EB), potential for safety improvement (PSI), and full Bayesian (FB) methods. To evaluate the performance of the HSID methods, hotspot consistency over two years was tested. The results showed 1) that EB and PSI performed better than the other methods no matter which research unit was used; 2) substantial inconsistency between the identified micro- and meso-level hotspots. To identify both hazardous corridors and individual intersections and road segments on urban arterials, a combination of micro- and meso-level hotspots should be recommended to local transportation authorities.

Detecting and Analyzing Mobility Hotspots using Surface Networks

Abstract:Capabilities for collecting and storing data on mobile objects have increased dramatically over the past few decades. A persistent difficulty is summarizing large collections of mobile objects. This paper develops methods for extracting and analyzing hotspots or locations with relatively high levels of mobility activity. We use kernel density estimation (KDE) to convert a large collection of mobile objects into a smooth, continuous surface. We then develop a topological algorithm to extract critical geometric features of the surface; these include critical points (peaks, pits and passes) and critical lines (ridgelines and course-lines). We connect the peaks and corresponding ridgelines to produce a surface network that summarizes the topological structure of the surface. We apply graph theoretic indices to analytically characterize the surface and its changes over time. To illustrate our approach, we apply the techniques to taxi cab data collected in Shanghai, China. We find increases in the complexity of the hotspot spatial distribution during normal activity hours in the late morning, afternoon and evening and a spike in the connectivity of the hotspot spatial distribution in the morning as taxis concentrate on servicing travel to work. These results match with scientific and anecdotal knowledge about human activity patterns in the study area.
