Abstract:Feedback-directed optimization (FDO) is effective in improving application runtime performance, but has not been widely adopted due to the tedious dual-compilation model, the difficulties in generating representative training data sets, and the high runtime overhead of profile collection. The use of hardware-event sampling overcomes these drawbacks by providing a lightweight approach to collect execution profiles in the production environment, which naturally consumes representative input. Yet, hardware event samples are typically not precise at the instruction or basic-block granularity. These inaccuracies lead to missed performance when compared to instrumentation-based FDO. In this paper, we use Performance Monitoring Unit (PMU)-based sampling to collect the instruction frequency profiles. By collecting profiles using multiple events, and applying heuristics to predict the accuracy, we improve the accuracy of the profile. We also show how emerging techniques can be used to further improve the accuracy of the sample-based profile. Additionally, these emerging techniques are used to collect value profiles, as well as to assist a lightweight interprocedural optimizer. All these profiles are represented in a portable form, thus they can be used across different platforms. We demonstrate that sampling-based FDO can achieve an average of 92 percent of the performance gains obtained using instrumentation-based exact profiles for both SPEC CINT2000 and CINT2006 benchmarks. The overhead of collection is only 0.93 percent on average, while compiler-based instrumentation incurs 2.0-351.5 percent overhead (and 10x overhead on an industrial web search application).

Abstract:Feedback-directed optimization (FDO) is effective in improving application runtime performance, but has not been widely adopted due to the tedious dual-compilation model, the difficulties in generating representative training data sets, and the high runtime overhead of profile collection. The use of hardware-event sampling to generate estimated edge profiles overcomes these drawbacks. Yet, hardware event samples are typically not precise at the instruction or basic-block granularity. These inaccuracies lead to missed performance when compared to instrumentation-based FDO@. In this paper, we use multiple hardware event profiles and supervised learning techniques to generate heuristics for improved precision of basic-block-level sample profiles, and to further improve the smoothing algorithms used to construct edge profiles. We demonstrate that sampling-based FDO can achieve an average of 78% of the performance gains obtained using instrumentation-based exact edge profiles for SPEC2000 benchmarks, matching or beating instrumentation-based FDO in many cases. The overhead of collection is only 0.74% on average, while compiler based instrumentation incurs 6.8%-53.5% overhead (and 10x overhead on an industrial web search application), and dynamic instrumentation incurs 28.6%-1639.2% overhead.

Abstract:A new compilation method with performance-optimized dynamic compound macro(PODCM)library was proposed for fast compilation of field programmable gate array(FPGA). After studying conditions for generating PODCM in the critical path of data flow graph(DFG),an algorithm was introduced to produce PODCM.Based on PODCM library and according to PODCM replacement algorithm,PODCMs were applied to replace nodes in the critical path of DFG,which provided significant reduction in DFG critical timing.Experiment results show that with high compilation speed and no increase of resources,the new compilation method can efficiently improve the performance of FPGA design.
A Sample Profile-Based Optimization Method with Better Precision

Abstract:Conventional feedback-directed optimization is not widely adopted for the difficulties in generating representative training data sets. High runtime overhead and tedious re-compilation model obstruct its usability. Instruction-level hardware event sampling may overcome the drawbacks. There are still several challenges in creating accurate edge profiles, which is necessary to achieve competitive performance gains. This paper focuses on multiple hardware event profiles, supervised learning to discover patterns and generate heuristics to improve the precision of the instruction-level sample profile. We further enhance the efficacy of the smoothing algorithm used to construct the edge profiles from the instruction level and basic-block level samples. With these improvements, it is able to achieve about 70% of the performance obtained via instrumentation-based exact edge profiles for SPEC benchmarks, which also brings better performance of about 2.05%-13.81% improvement.
A Dynamic Resource Allocation Optimization for SMT Processors

Abstract:The threads on simultaneous multithreading (SMT) processors compete for the common resources rather than share them, and meanwhile they take on changing program phases. It is a challenge to meet the changing resource requirements of the threads by making resource allocation according to limited pipeline information. To avoid the stagnation of resource allocation optimization in the local suboptimal resource distributions and perform quick capture on the new optimal resource distributions, this paper proposes a dynamic resource allocation optimization (DRAO) for SMT processors, which optimizes the resource allocation targeting only the throughput performance. An optimization model with consideration of both throughput and fairness performance is designed for DRAO to steer the exploitation on historical allocation and the exploration on new allocation solutions. Results from experiment show that DRAO obtains potential improvement of fairness performance as well as good improvement of throughput performance. These are attributed to the well-balanced exploitation and exploration activities.
FADO: Floorplan-Aware Directive Optimization for High-Level Synthesis Designs on Multi-Die FPGAs

Abstract:Multi-die FPGAs are widely adopted to deploy large hardware accelerators. Two factors impede the performance optimization of HLS designs implemented on multi-die FPGAs. On the one hand, the long net delay due to nets crossing die-boundaries results in an NP-hard problem to properly floorplan and pipeline an application. On the other hand, traditional automated searching flow for HLS directive optimizations targets single-die FPGAs, and hence, it cannot consider the resource constraints on each die and the timing issue incurred by the die-crossings. Further, it leads to an excessively long runtime to legalize the floorplan of HLS designs generated under each group of configurations during directive optimization due to the large design scale. To co-optimize the directives and floorplan of HLS designs on multi-die FPGAs, we propose the FADO framework, which formulates the directive-floorplan co-search problem based on the multi-choice multi-dimensional bin-packing and solves it using an iterative optimization flow. For each step of directive search, a latency-bottleneck-guided greedy algorithm searches for more efficient directive configurations. For floorplanning, instead of repetitively incurring global floorplanning algorithms, we implement a more efficient incremental floorplan legalization algorithm. It mainly applies the worst-fit online bin-packing algorithm to balance the floorplan, together with an offline best-fit-decreasing re-packing to compact the floorplan, followed by pipelining of long wires crossing die-boundaries. Through experiments on HLS designs mixing dataflow and non-dataflow kernels, FADO not only well-automates the co-optimization and finishes within 693X~4925X shorter runtime, compared with DSE assisted by global floorplanning, but also yields an improvement of 1.16X~8.78X in overall workflow execution time after implementation on the Xilinx Alveo U250 FPGA.

Abstract:The optimization of the application of complex scientific computation was studied to face the challenge that the complexity of high performance computers grows quickly with their performance increasing, and the CPTF, a hardware/software co design performance tuning framework, was proposed. The CPTF can give an overall analysis of a computer system’s performance bottlenecks and their types according to the profile of the application at run time combined with the application’s software characters and the platform’s hardware characters, and finally give optimization suggestions on source level. And also it can propose an advanced loop fusion algorithm to solve the common problems in loop optimizing. The CPTF was used to optimize the particles simulation application of MPM and achieved about 20% of performance improvement.

Abstract:Multi-die FPGAs are widely adopted for large-scale accelerators, but optimizing high-level synthesis designs on these FPGAs faces two challenges. First, the delay caused by die-crossing nets creates an NP-hard floorplanning problem. Second, traditional directive optimization cannot consider resource constraints on each die or the timing issue incurred by the die-crossings. Furthermore, the high algorithmic complexity and the large scale lead to extended runtime for legalizing the floorplan of HLS designs under different directive configurations. To co-optimize the directives and floorplan of HLS designs on multi-die FPGAs, we formulate the co-search based on bin-packing variants and present two iterative optimization flows. The first (FADO 1.0) relies on a pre-built QoR library. It involves a greedy, latency-bottleneck-guided directive search and an incremental floorplan legalization. Compared with a global floorplanning solution, it takes 693X ∼ 4925X shorter search time and achieves 1.16X ∼ 8.78X better design performance, measured in workload execution time. To remove the time-consuming QoR library generation, the second flow (FADO 2.0) integrates an analytical QoR model and redesigns the directive search to accelerate convergence. Through experiments on mixed dataflow and non-dataflow designs, compared with 1.0, FADO 2.0 further yields a 1.40X better design performance on average after implementation on the Alveo U250 FPGA.

Abstract:Progress in co-processor acceleration has enabled fast and high-performance deployment of intensive computation applications such as deep learning algorithms. Recently, new heterogeneous cooperation patterns have been studied to produce further acceleration on discrete or large-scale computing systems. Hence, in this paper, we explore auto-tuning strategies for task scheduling in heterogeneous cooperation between kernel operators. The tuning outcomes are designed to work in harmony with the kernel operators optimized by the TVM compiler. To hook up with the mainstream frameworks, we build a toolchain based on the Heterogeneous System Architecture (HSA) and the ROCM platform for deep learning deployment. Compared with the original TVM and official TensorFlow on the ROCM platform, our work achieves a higher inference speed.
Feedback Scheduling of Real-Time Control Tasks in Power-Aware Embedded Systems

Abstract:Power awareness has become a critical issue in real-time scheduling of embedded systems. In the context of control applications, the goal of high control performance and low energy consumption are at odds with each other. While dynamic voltage/frequency scaling (DVS) has proved to be promising in energy saving while preserving task schedulability, traditional DVS algorithms use either open loop or ad hoc solutions, and hence cannot perform well for dynamic systems where the workload varies significantly. By targeting these systems, a novel scheme, namely DVS-FS, which combines DVS and feedback scheduling, is suggested. The objective is to save CPU energy as much as possible, while still providing control performance guarantees, which largely depends on successful schedule of the control task set. DVS-FS exploits feedback control methodology, and facilitates tradeoffs between energy consumption and control performance through controlling the CPU utilization at a considerably high level. Simulation experiments demonstrate that DVS-FS can easily reduce significant energy consumption at the expense of only minor control performance degradation.

Abstract:The performance of multitasking control systems with resource constraints depends not only on controller design, but also on efficient scheduling of the shared computing resources. To sup- port codesign of feedback control and real-time scheduling under overload conditions, a direct feedback scheduling approach is proposed. The goal is to optimize the overall system perform- ance through dynamically allocating limited CPU time based on control requirements. A con- trol application oriented task model is suggested, providing an interface between control per- formance and task scheduling decision. Abstract:Manual engineering of high-performance implementations typically consumes many resources and requires in-depth knowledge of the hardware. Compilers try to address these problems; however, they are limited by design in what they can do. To address this, we present CryptOpt, an automatic optimizer for long stretches of straightline code. Experimental results across eight hardware platforms show that CryptOpt achieves a speed-up factor of up to 2.56 over current off-the-shelf compilers.

Taming the "Monster": Overcoming Program Optimization Challenges on SW26010 Through Precise Performance Modeling

Abstract:This paper presents an effort for overcoming the complexities of program optimizations on SW26010, the heterogeneous many-core processor that powers Sunway TaihuLight, the world top one supercomputer. The solution centers around a precise, static performance model for modern many-core processor. Through a careful design that leverages the special properties of SW26010 and an effective treatment to massive parallelism, the model achieves a high accuracy, showing less than 5% average errors in estimating program execution performance. The precise performance model opens many opportunities for analyzing and guiding code optimizations. The paper demonstrates the usefulness by revealing a series of insights on the effects of some important code optimizations on SW26010. Moreover, it demonstrates that with such a precise performance model, it is feasible to replace empirical auto-tuning with static auto-tuning for optimizing regular loops on heterogeneous many-core systems. Such a replacement speeds up the tuning process by as much as a factor of 43 while keeping the tuning quality loss below 6%.

Abstract:Many applications, such as medical imaging, generate intensive data traffic between the FPGA and off-chip memory. Significant improvements in the execution time can be achieved with effective utilization of on-chip (scratchpad) memories, associated with careful software-based data reuse and communication scheduling techniques. We present a fully automated C-to-FPGA framework to address this problem. Our framework effectively implements data reuse through aggressive loop transformation-based program restructuring. In addition, our proposed framework automatically implements critical optimizations for performance such as task-level parallelization, loop pipelining, and data prefetching. We leverage the power and expressiveness of the polyhedral compilation model to develop a multi-objective optimization system for off-chip communications management. Our technique can satisfy hardware resource constraints (scratchpad size) while still aggressively exploiting data reuse. Our approach can also be used to reduce the on-chip buffer size subject to bandwidth constraint. We also implement a fast design space exploration technique for effective optimization of program performance using the Xilinx high-level synthesis tool.

Abstract:Mainstream FPGA tools contain an extensive set of user-controlled compilation options and internal optimization strategies that significantly impact the design quality. These compilation and optimization parameters create a complex design space that human designers may not be able to effectively explore in a time-efficient manner. In this work we describe DATuner, an open-source extensible distributed autotuning framework for optimizing FPGA designs and design automation tools using an ensemble of search techniques managed by multi-armed bandit algorithms. DATuner is designed for a distributed environment that uses parallel searches to amortize the significant runtime overhead of the CAD tools. DATuner provides convenient interface for extension to user-supplied tools, which enables the end users to apply DATuner to design tools/flows of their interest. We demonstrate the effectiveness and extensibility of DATuner using three case studies, which include clock frequency optimization for FPGA compilation, fixed-point optimization, and autotuning logic synthesis transformations.
ACC Saturator: Automatic Kernel Optimization for Directive-Based GPU Code

Abstract:Automatic code optimization is a complex process that typically involves the application of multiple discrete algorithms that modify the program structure irreversibly. However, the design of these algorithms is often monolithic, and they require repetitive implementation to perform similar analyses due to the lack of cooperation. To address this issue, modern optimization techniques, such as equality saturation, allow for exhaustive term rewriting at various levels of inputs, thereby simplifying compiler design. In this paper, we propose equality saturation to optimize sequential codes utilized in directive-based programming for GPUs. Our approach realizes less computation, less memory access, and high memory throughput simultaneously. Our fully-automated framework constructs single-assignment forms from inputs to be entirely rewritten while keeping dependencies and extracts optimal cases. Through practical benchmarks, we demonstrate a significant performance improvement on several compilers. Furthermore, we highlight the advantages of computational reordering and emphasize the significance of memory-access order for modern GPUs.

3-Regular 3-XORSAT Planted Solutions Benchmark of Classical and Quantum Heuristic Optimizers

Abstract:With current semiconductor technology reaching its physical limits, special-purpose hardware has emerged as an option to tackle specific computing-intensive challenges. Optimization in the form of solving Quadratic Unconstrained Binary Optimization (QUBO) problems, or equivalently Ising spin glasses, has been the focus of several new dedicated hardware platforms. These platforms come in many different flavors, from highly-efficient hardware implementations on digital-logic of established algorithms to proposals of analog hardware implementing new algorithms. In this work, we use a mapping of a specific class of linear equations whose solutions can be found efficiently, to a hard constraint satisfaction problem (3-regular 3-XORSAT, or an Ising spin glass) with a 'golf-course' shaped energy landscape, to benchmark several of these different approaches. We perform a scaling and prefactor analysis of the performance of Fujitsu's Digital Annealer Unit (DAU), the D-Wave Advantage quantum annealer, a Virtual MemComputing Machine, Toshiba's Simulated Bifurcation Machine (SBM), the SATonGPU algorithm from Bernaschi et al., and our implementation of parallel tempering. We identify the SATonGPU and DAU as currently having the smallest scaling exponent for this benchmark, with SATonGPU having a small scaling advantage and in addition having by far the smallest prefactor thanks to its use of massive parallelism. Our work provides an objective assessment and a snapshot of the promise and limitations of dedicated optimization hardware relative to a particular class of optimization problems.

An Experience-Guided Acceleration Strategy for Floating-Point Optimization

Abstract:To ensure the correctness and efficiency of floating-point programs, automatic optimizing techniques for floating-point programs have been attached attention from academia in recent years. The core idea is to summarize transformation rules from classical numerical analysis theory and rewrite floating-point programs automatically with more stable algorithms, which produces more stable, efficient and maintainable programs. However, efficiency becomes the bottleneck of these techniques. As more and more transformation rules are discovered and summarized, the rule base used by the optimizing framework becomes larger and larger. It is more difficult to scan the whole rule base as usual. In this paper, we propose an experience-guided acceleration strategy for floatingpoint optimization. Based on the principle of similar causes of floating-point errors, the strategy extracts the corresponding symbolic and structural features of successfully optimized floating-point programs, and saves the rule sequences involved in the optimization of the programs into a hash-based optimization experience database. When optimizing a floating-point program, the optimizer first calculates the similarity between symbolic and structural features of the program and that of records in the experience base. Rule sequences associated with records having higher similarity are preferred to be used in rewriting and optimizing the program. With more and more programs to be optimized, the experience base increases gradually and a hashed-partition design ensures the efficiency of record-searching. The above approach has been evaluated on the FPBench benchmark and the open source engine OpenRelativity. The results show that compared to the traditional optimizing approach, it can achieve a 6.04x speedup in average. In addition, it improves accuracy for floating-point programs effectively as well as the traditional optimizing approach does. Therefore, our approach improves the usability of automatic optimizing techniques significantly.
A Comprehensive Methodology to Optimize FPGA Designs via the Roofline Model

Abstract:With reconfigurable fabrics delivering increasing performance over the years, Field-Programmable Gate Arrays (FPGAs) are becoming an appealing solution for next-generation High-Performance Computing (HPC) systems. However, in order to gain traction among traditional von Neumann architectures, the optimization process of Field-Programmable Gate Array (FPGA) designs should be further abstracted to a higher level. In fact, while High-Level Synthesis (HLS) already provides a handy way to write FPGA code with common high-level languages, substantial effort and expertise are still required to optimize the resulting FPGA design for the underlying hardware. To overcome this problem, we propose a semi-automated performance optimization methodology based on a Hierarchical Roofline model for FPGAs. System-wide and applications-specific optimizations such as off-chip memory transfer and data locality optimizations are guided by the FPGA Roofline model whereas FPGA-specific optimizations are automatically searched by a Design Space Exploration (DSE) engine. We demonstrate the way this methodology allows to easily analyze and optimize to peak system performance a wide set of applications ranging from particle methods, wavefront algorithms, and sparse arithmetic computations. In addition, we prove that the integrated Design Space Exploration (DSE) engine achieves a 14.36x maximum speedup if compared to previous automated solutions in the literature.

Abstract:The accuracy of debugging information is crucial for source level debugging. However the debugging information may be inaccurate after sophisticated optimizations if the target program is compiled into native code. Hence, the efficiency of diagnosing software is affected due to inaccurate debugging information. To address the issue, we propose Debugopt, a framework for debugging fully optimized natively compiled programs using multistage instrumentation. At compile time, Debugopt generates unoptimized programs with accurate debugging information and optimized programs. At debugging time, Debugopt dynamically replaces the execution of optimized programs with unoptimized programs. Debugopt is implemented on multiple architectures, including x86-32, x86-64, armv7 and mips3. Debugopt's overhead is small during normal execution on a large range of benchmarks.
