Abstract:Poor road conditions are a public nuisance, causing passenger discomfort, damage to vehicles, and accidents. In the U.S., road-related conditions are a factor in 22,000 of the 42,000 traffic fatalities each year. Although we often complain about bad roads, we have no way to detect or report them at scale. To address this issue, we developed a system to detect potholes and assess road conditions in real-time. Our solution is a mobile application that captures data on a car's movement from gyroscope and accelerometer sensors in the phone. To assess roads using this sensor data, we trained SVM models to classify road conditions with 93% accuracy and potholes with 92% accuracy, beating the base rate for both problems. As the user drives, the models use the sensor data to classify whether the road is good or bad, and whether it contains potholes. Then, the classification results are used to create data-rich maps that illustrate road conditions across the city. Our system will empower civic officials to identify and repair damaged roads which inconvenience passengers and cause accidents. This paper details our data science process for collecting training data on real roads, transforming noisy sensor data into useful signals, training and evaluating machine learning models, and deploying those models to production through a real-time classification app. It also highlights how cities can use our system to crowdsource data and deliver road repair resources to areas in need.

Abstract:Identifying and fixing roadway potholes promptly can improve roadway safety and decrease vehicular damage, which is essential in transportation infrastructure management. Transportation agencies are constantly looking for efficient solutions for pavement intelligent management and maintenance. Traditionally, laser scanning, accelerometers, and videos are the major detecting sources employed to diagnose pavement distress. However, the responsiveness of these methods is constrained by the limited amount of equipment and labor. By contrast, popular crowdsourced tools like the navigation app Waze provide citizens with a cost-effective way to feed real-time roadway information, which could facilitate the evaluation, detection, and repair of potholes. To examine these possibilities, the study collected one-year pothole reports for five critical corridors in Nashville, Tennessee as a case study. Firstly, a Spatial Temporal Kernel Density Estimation (STKDE) was proposed to estimate the likelihood of potholes over space and time. The results highlight the spatiotemporal variation of pothole propensity. Furthermore, the hotspots recognized at a 95% confidence level revealed the significantly vulnerable areas and times, such as I-40 Westbound near log mile marker 13 from January to June 2021. Secondly, based on the optimal bandwidths generated by STKDE, spatiotemporal DBSCAN clustering was performed to identify potholes. Two pothole patterns are identified and interpreted as isolated spots and pothole zones, respectively. It was also found that crowdsourced reports come up much sooner than work requests in the Pavement Management System (PMS). Moreover, pothole reports also identified several blind spots ignored by the maintenance team. This study contributes to facilitating pavement management and maintenance with emerging crowdsourced data.

Abstract:Road conditions with holes are a common cause of accidents in a traffic environment. For motorcycle riders, car drivers, and other vehicle drivers, this can be fatal. For driving comfort, transportation safety, and infrastructure integrity, road surface monitoring and maintenance are critical. As a result, by identifying pot holes on the highway, this article seeks to develop a road contour damage information system. In this work, we suggest an Android-based application for executing data collecting points for government entities such as the NHAI and municipalities, among others. To create the app, we trained a model to recognize whether or not an image has a pothole. If a pothole is detected, the image is saved on a server, where it can subsequently be retrieved by appropriate authorities for maintenance and analysis. Instead of using the classic paper pen method, government personnel can utilise this mobile app to collect data. We plan to limit the quantity of photographs a person can upload because data can be very large. The findings of this study are expected to play a significant role in guaranteeing safe driving in the future by effectively detecting poor road conditions.
YOLOv5-Pothole: an Improved Pothole Perception Method Based on YOLOv5-Seg

Abstract:Road pothole damage represents a significant challenge in transportation infrastructure. Numerous studies have aimed to automate pothole detection by employing diverse computer vision techniques. There is a critical need for an automated road pothole detection process that offers sufficient accuracy and speed, while also being cost-effective and straightforward to implement. We introduce an enhanced road pothole detection algorithm, YOLOv5-pothole, based on the YOLOv5-seg model. Inputs for this algorithm include RGB images, depth images, and camera position data, all captured by a D455 depth camera. Concurrently, LiDAR sensors are used to acquire 3D point cloud data. The RGB images are semantically segmented by the self-trained YOLOv5-seg network, and corresponding virtual point clouds are generated through coordinate transformation. Then we register the 3D point clouds with the virtual point clouds generated from 2D pothole images to supplement the semantic information of the pothole. Finally, the pothole point clouds are individually segmented using Euclidean clustering, providing the information of the pothole. The GRDDC2020 experimental dataset was used to train the YOLOv5-seg network. We tested the YOLOv5-pothole algorithm on five randomly selected road potholes, with experimental results indicating a mean detection error of 7.0%. The algorithm demonstrated effective detection across potholes of varying sizes. This study offers valuable insights for future real-time road pothole detection research.

Abstract:In developing countries, road maintenance is a major problem. The country's economy relies significantly on public transit. Driving a vehicle on a badly maintained road is very dangerous. Rain causes the road's oil-spill quality to degrade. Car accidents may occur as a result of such obstacles. To solve this problem, we have developed a project that we believe would be of the most use to the public. The project's main aim is to automatically detect and report potholes. This article discusses a cost-effective method for detecting potholes and speed bumps on roadways, as well as giving timely warnings to drivers to assist them avoid accidents or vehicle damage. Potholes and humps are detected using ultrasonic sensors, which may also be utilised to assess their depth and height. A global positioning system receiver is used in the proposed system to record the geographic locations of potholes and speed bumps. Some of the discovered data in the database include pothole depth, hump height, and geographic location. This is a valuable resource for both government officials and motorists. As an alert, flash messages with an audible buzzer are used.

Abstract:Real-time road quality monitoring, involves using technologies to collect data on the conditions of the road, including information on potholes, cracks, and other defects. This information can help to improve safety for drivers and reduce costs associated with road damage. Traditional methods are time-consuming and expensive, leading to limited spatial coverage and delayed responses to road conditions. With the widespread use of smartphones and ubiquitous computing technologies, data can be collected from built-in sensors of mobile phones and in-vehicle video, on a large scale. This has raised the question of how these data can be used for road pothole detection and has significant practical relevance. Current methods either use acceleration sequence classification techniques, or image recognition techniques based on deep learning. However, accelerometer-based detection has limited coverage and is sensitive to the driving speed, while image recognition-based detection is highly affected by ambient light. To address these issues, this study proposes a method that utilizes the fusion of accelerometer data and in-vehicle video data, which is uploaded by the participating users. The preprocessed accelerometer data and intercepted video frames, were then encoded into real-valued vectors, and projected into the public space. A deep learning-based training approach was used to learn from the public space and identify road anomalies. Spatial density-based clustering was implemented in a multi-vehicle scenario, to improve reliability and optimize detection results. The performance of the model is evaluated with confusion matrix-based classification metrics. Real-world vehicle experiments are carried out, and the results demonstrate that the proposed method can improve accuracy by 6% compared to the traditional method. Consequently, the proposed method provides a novel approach for large-scale pavement anomaly detection.

Abstract:This paper presents a VIDAR (a Vision-IMU based detection and ranging method)-based approach to road-surface pothole detection. Most potholes on the road surface are caused by the further erosion of cracks in the road surface, and tires, wheels and bearings of vehicles are damaged to some extent as they pass through the potholes. To ensure the safety and stability of vehicle driving, we propose a VIDAR-based pothole-detection method. The method combines vision with IMU to filter, mark and frame potholes on flat pavements using MSER to calculate the width, length and depth of potholes. By comparing it with the classical method and using the confusion matrix to judge the correctness, recall and accuracy of the method proposed in this paper, it is verified that the method proposed in this paper can improve the accuracy of monocular vision in detecting potholes in road surfaces.

Abstract:Road infrastructure degradation remains a significant challenge, prompting the utilization of cutting-edge image processing techniques to enhance infrastructure management and road safety. While traditional pothole patching methods are time-consuming, this research study focuses on three key aspects of road maintenance: assessing the prevalence of potholes, evaluating their impact on road conditions, and alerting drivers to nearby potholes to mitigate risks. To differentiate from approaches that merely detect and count potholes, the proposed methodology incorporates segmentation techniques to precisely quantify areas impacted by potholes. This involves utilizing the capabilities of a YOLOv8 model trained on custom real-time image datasets. The YOLOv8 model stands out for its user-friendly interface, simplicity, and effectiveness, as highlighted in this research. Moreover, this study introduces a novel route selection method based on the severity of road damage and pothole presence. The main aim of this study is to substantially enhance road safety, refine maintenance practices, and reinforce the resilience of urban environments through these innovative solutions.

Abstract:Road discrepancies such as potholes and road cracks are often present in our day-to-day commuting and travel. The cost of damage repairs caused by potholes has always been a concern for owners of any type of vehicle. Thus, an early detection processes can contribute to the swift response of road maintenance services and the prevention of pothole related accidents. In this paper, automatic detection of potholes is performed using the computer vision model library, You Look Only Once version 3, also known as Yolo v3. Light and weather during driving naturally affect our ability to observe road damage. Such adverse conditions also negatively influence the performance of visual object detectors. The aim of this work was to examine the effect adverse conditions have on pothole detection. The basic design of this study is therefore composed of two main parts: (1) dataset creation and data processing, and (2) dataset experiments using Yolo v3. Additionally, Sparse R-CNN was incorporated into our experiments. For this purpose, a dataset consisting of subsets of images recorded under different light and weather was developed. To the best of our knowledge, there exists no detailed analysis of pothole detection performance under adverse conditions. Despite the existence of newer libraries, Yolo v3 is still a competitive architecture that provides good results with lower hardware requirements.

Abstract:Traditional pothole detection based on two-dimensional images lacks three-dimensional (3D) quantitative information such as depth and volume, although the high accuracy. In addition, existing 3D collection and reconstruction equipment based on depth cameras and lasers are expensive and difficult to operate. To solve the above problems, a low cost and automatic 3D reconstruction and segmentation system for potholes is proposed in this study. The system consists of a pavement pothole Structure-from-motion (PP-SFM) and a 3D point cloud segmentation network for potholes. Firstly, a point cloud reconstruction method called PP-SFM is proposed to reconstruct the easily obtained multi-view 2D potholes images. In addition, to a certain extent, the point cloud sparse problem is solved by the proposed PP-SFM, and the stereo display of potholes is realized. Next, Trans-3D-Seg is developed based on an improved 3D segmentation network modified by the transformer module to ealize effective segmentation of 3D point cloud data of potholes. The accuracy of the improved system is 93.44%, and the F1-score is 92.58%. In addition, the precision-recall (P-R) curve is near the upper right. Comparative experiments show that the proposed system has better segmentation performance. Compared with PointNet++, PointRCNN and PointCNN, the segmentation accuracy are increased by 4.13%, 2.96% and 3.17%, respectively. The F1-score are increased by 2.41%, 2.43% and 2.93%, respectively. The proposed system requires only a few multi-view images taken from ordinary high-definition cameras, which is a high accuracy and low cost method for 3D reconstruction and segmentation of pavement potholes.

Abstract:In this paper, we propose a centralized system which detects potholes on roads and assists the driver to avoid them. The system consists of 3 components namely sensors for detection, an inter-vehicle communication protocol to warn other vehicles about the new potholes which are detected, a central server which maintains a database of all the potholes. The system also consists of a GPS navigation system which will route the vehicle through an efficient path based on certain paramaters such as length of the route, intensity of potholes in the route, vehicle load and type, size limits of the road etc. In addition to this, the central server is configured to assign priority to the potholes and report high priority potholes to any local council such as a municipality so that they are repaired immediately.

Abstract:Potholes are a serious issue with the road network that endangers drivers' safety and seriously damages cars. Timely repairs and upkeep of roads depend on the accurate and real-time identification of potholes. Numerous studies have b een conducted on pothole identification among other pavement problems since they can cause injuries to cars and passengers and result in an accident. The research study explores how potholes can be detected using deep learning (DL. The study depends mainly on the well-known (You Look Only Once) YOLO model, examined on a Publicly available dataset from Kaggle, For Efficient detection of potholes canny edge detection techniques are also used to enhance the model accuracy. The research depicts that the YOLOv8 model is very effective when it comes to finding potholes as it has an accuracy of 99.2%. The results show that the issue of potholes can be detected and fixed using YOLOv8 in a way where the road is safe for everyone.

Abstract:To propose a single-stage object detection method for realizing realtime and accurate identification and detection of near-ground small pothole objects photographed by UAV. Through the special copy-paste technology of the pothole dataset obtained by the drone, combined with the key point detection branch, the Anchor and loss function are redesigned and improving the Soft-NMS. The automatic detection of near-ground small objects is finally realized. Results: On the pothole data set, the detection of the 4000 * 3000 size map can be completed within 6 s, and theAP on the test set can reach 85%. The experimental results show that the algorithm can not only accurately identify the potholes in the near-ground roads, but also meet the real-time requirements, and can be deployed on UAVs to detect near-ground objects such as potholes.

Abstract:Automatic detection and rapid extraction of condition characteristics of pavement potholes are important support for road health monitoring and maintenance. In this paper, a method of extracting pavement potholes in vehicle-borne continuous laser point cloud combined with two-dimensional and three-dimensional analysis is proposed. This method mainly includes three parts: Firstly, point cloud data preprocessing is carried out to remove non-road point cloud and road noise points; Then the transverse and longitudinal sections of the road are extracted according to the scanning line index of the laser point cloud. The Douglas-Pucker operator is used to analyse the profile contour characteristics, and the integral invariant operator is used to identify the initial feature points of the pothole; Finally, the local datum surface of the pavement is constructed by fitting, and the continuous depth image of the pavement is generated. The active contour model operator is used to accurately extract the pothole boundary based on the local depth information, and the geometric information such as the depth and area of the pothole is obtained. Select some road point cloud data for experiments, the results show that the pothole feature point extraction method in this paper is relatively robust, the extraction precision rate reaches 86.1%, and the recall rate reaches 91.2%. By generating a local depth image for precise extraction of the pothole boundary, it can effectively solve the problem of inaccurate extraction of the pothole boundary based on discrete point clouds. Compared with the manual measurement results, the relative error of the area is less than 7%, and the relative error of the depth is less than 6%, which proves the effectiveness of this method.

Abstract:Abstract Today, the number of vehicles using the road including highways and single carriage way is increasing. road structure safety monitoring system that is safe for road users and also important to ensure long-term vehicle safety and prevent accidents due to road damage such as potholes, landslides and uneven roads. Most news reports of road accidents are also caused by potholes that are almost 10-30 cm deep, coupled with heavy rainfall that reduces visibility among drivers, significant damage to the suspension system to the vehicle or unnecessary traffic congestion. In this paper, deep learning detection with YOLOv3 algorithm is proposed apart from researches ranging from accelerometer detection, image processing or machine learning based detection as it is easier to develop and provide more accurate results. After pothole has been detected in real-time webcam, the location will be logged and displayed using Google Maps API for visualization. a total of 330 sets of data were sampled for the implementation of the pothole detection training model. As the results, the model provided 65.05 mAP and 0.9 % precision rate and 0.41 recall rate. The limitation of YOLOv3 algorithm detection can be improve further using GPU with higher specification performances and can sample 1000 to 10,000 datasets. The proposed algorithm provides acceptably high precision and efficient pothole monitoring solution under different scenarios for the users and may benefit the public and the government to monitor pothole in real-time.
An Automated Machine-Learning Approach for Road Pothole Detection Using Smartphone Sensor Data

Abstract:Road surface monitoring and maintenance are essential for driving comfort, transport safety and preserving infrastructure integrity. Traditional road condition monitoring is regularly conducted by specially designed instrumented vehicles, which requires time and money and is only able to cover a limited proportion of the road network. In light of the ubiquitous use of smartphones, this paper proposes an automatic pothole detection system utilizing the built-in vibration sensors and global positioning system receivers in smartphones. We collected road condition data in a city using dedicated vehicles and smartphones with a purpose-built mobile application designed for this study. A series of processing methods were applied to the collected data, and features from different frequency domains were extracted, along with various machine-learning classifiers. The results indicated that features from the time and frequency domains outperformed other features for identifying potholes. Among the classifiers tested, the Random Forest method exhibited the best classification performance for potholes, with a precision of 88.5% and recall of 75%. Finally, we validated the proposed method using datasets generated from different road types and examined its universality and robustness.

Abstract:In the field of computer vision, the detection of road potholes at night represents a critical challenge in enhancing the safety of intelligent transportation systems. Ensuring road safety is of paramount importance, particularly in promptly repairing pothole issues. These abrupt road depressions can easily lead to vehicle skidding, loss of control, and even traffic accidents, especially when water has pooled in or submerged the potholes. Therefore, the detection and recognition of road potholes can significantly reduce vehicle damage and the incidence of safety incidents. However, research on road pothole detection lacks high-quality annotated datasets, particularly under low-light conditions at night. To address this issue, this study introduces a novel Nighttime Pothole Dataset (NPD), independently collected and comprising 3831 images that capture diverse scene variations. The construction of this dataset aims to counteract the insufficiency of existing data resources and strives to provide a richer and more realistic benchmark. Additionally, we develop a baseline detector, termed WT-YOLOv8, for the proposed dataset, based on YOLOv8. We also evaluate the performance of the improved WT-YOLOv8 method and eight state-of-the-art object detection methods on the NPD and the COCO dataset. The experimental results on the NPD demonstrate that WT-YOLOv8 achieves a 2.3% improvement in mean Average Precision (mAP) over YOLOv8. In terms of the key metrics—AP@0.5 and AP@0.75—it shows enhancements of 1.5% and 2.8%, respectively, compared to YOLOv8. The experimental results provide valuable insights into each method's strengths and weaknesses under low-light conditions. This analysis highlights the importance of a specialized dataset for nighttime pothole detection and shows variations in accuracy and robustness among methods, emphasizing the need for improved nighttime pothole detection techniques. The introduction of the NPD is expected to stimulate further research, encouraging the development of advanced algorithms for nighttime pothole detection, ultimately leading to more flexible and reliable road maintenance and road safety.

Abstract:Automated detection of pavement distress can prevent deterioration of premature surface disintegration in pavements. Potholes that are a common sight in harsh and cold terrains are a severe threat to road safety and a major contributing factor to pavement distress. To facilitate timely detection and repair of potholes, a computationally light and feasible, intelligent pavement pothole detection system is proposed by developing a novel workflow for image-based detection and severity assessment. A single-stage CNN architecture, RetinaNet is modified and optimised to best detect potholes and used in combination with a novel pothole depth estimation algorithm. A comparative evaluation of the model's performance against the existing state-of-the-art model on the benchmark dataset establishes the proposed model's high performance and applicability in real-time scenarios. The depth estimation algorithm is based on a 3D road surface model generated by employing the photogrammetric process of structure from motion (SfM). The point cloud data obtained thereafter, is used for accurate measurement of pothole depth. The comparison of the derived depth with the onsite depth measurement of the pothole reveals a mean error below 5%. This method leads to a practical and intelligent solution to be implemented as part of a potential pavement health assessment system for future practice.

A Modified Pothole Detection Approach to Capture their Width

Abstract:Detecting potholes is an ongoing problem that requires extensive investigations as potholes significantly deteriorate urban beauty and can cause serious harm to commuters. Multiple techniques have been developed over the years to address that issue. However, there has been no formal way to define the size, particularly the width, of a pothole. This work presents a mathematical definition for the width of an arbitrary 2D pothole at a point inside. Then, the width of each pothole is calculated by taking the supremum of all width values at all points in a given subset of that pothole. We also extend the detection pipeline by Koch and Brilakis in 2011 to prove the practicality of these definitions. The obtained experimental results show that our modification improves the pothole segmentation. Consequently, it gives a more accurate estimation of pothole widths.
