Abstract:Inspired by the observation that a healthcare system usually involves various intelligent technologies from different disciplines, especially metaheuristics and data mining, this paper provides a brief survey of metaheuristics for healthcare system and a roadmap for researchers working on metaheuristics and healthcare to develop a more efficient and effective healthcare system. This paper begins with a discussion of changes for healthcare, followed by a brief review of the features of "up-to-date technologies for healthcare.". Then, a learnable big data analytics framework for healthcare system is presented which provides a high performance solution to the forthcoming challenges of big data. Finally, changes, potentials, open issues, and future trends of metaheuristics for healthcare are addressed. (C) 2016 Elsevier Ltd. All rights reserved.

Abstract:Metaheuristic algorithms have emerged in recent years as effective computational tools for addressing complex optimization problems in many areas, including healthcare. These algorithms can efficiently search through large solution spaces and locate optimal or near-optimal responses to complex issues. Although metaheuristic algorithms are crucial, previous review studies have not thoroughly investigated their applications in key healthcare areas such as clinical diagnosis and monitoring, medical imaging and processing, healthcare operations and management, as well as public health and emergency response. Numerous studies also failed to highlight the common challenges faced by metaheuristics in these areas. This review thus offers a comprehensive understanding of metaheuristic algorithms in these domains, along with their challenges and future development. It focuses on specific challenges associated with data quality and quantity, privacy and security, the complexity of high-dimensional spaces, and interpretability. We also investigate the capacity of metaheuristics to tackle and mitigate these challenges efficiently. Metaheuristic algorithms have significantly contributed to clinical decision-making by optimizing treatment plans and resource allocation and improving patient outcomes, as demonstrated in the literature. Nevertheless, the improper utilization of metaheuristic algorithms may give rise to various complications within medicine and healthcare despite their numerous benefits. Primary concerns comprise the complexity of the algorithms employed, the challenge in understanding the outcomes, and ethical considerations concerning data confidentiality and the well-being of patients. Advanced metaheuristic algorithms can optimize the scheduling of maintenance for medical equipment, minimizing operational downtime and ensuring continuous access to critical resources.

Abstract:As a subset of machine learning, meta-learning, or learning to learn, aims at improving the model's capabilities by employing prior knowledge and experience. A meta-learning paradigm can appropriately tackle the conventional challenges of traditional learning approaches, such as insufficient number of samples, domain shifts, and generalization. These unique characteristics position meta-learning as a suitable choice for developing influential solutions in various healthcare contexts, where the available data is often insufficient, and the data collection methodologies are different. This survey discusses meta-learning broad applications in the healthcare domain to provide insight into how and where it can address critical healthcare challenges. We first describe the theoretical foundations and pivotal methods of meta-learning. We then divide the employed meta-learning approaches in the healthcare domain into two main categories of multi/single-task learning and many/few-shot learning and survey the studies. Finally, we highlight the current challenges in meta-learning research, discuss the potential solutions, and provide future perspectives on meta-learning in healthcare.

Abstract:Accurate and rapid disease detection is necessary to manage health problems early. Rapid increases in data amount and dimensionality caused challenges in many disciplines, with the primary issues being high computing costs, memory costs, and low accuracy performance. These issues will arise since Machine Learning (ML) classifiers are mostly used in these fields. However, noisy and irrelevant features have an impact on ML accuracy. Therefore, to choose the best subset of features and decrease the dimensionality of the data, Metaheuristics (MHs) optimization algorithms are applied to Feature Selection (FS) using various modalities of medical imaging or disease datasets with different dimensions. The review starts by giving a general overview of the many approaches to AI algorithms, followed by a general overview of the various MH algorithms for healthcare applications, an analysis of MHs boosted AI for healthcare applications, and using a wide range of research databases as a data source for access to numerous field publications. The final section of this review discusses the problems and challenges facing healthcare application development.

Abstract:In recent years vast quantities of data have been managed in various ways of medical applications and multiple organizations worldwide have developed this type of data and, together, these heterogeneous data are called big data. Data with other characteristics, quantity, speed and variety are the word big data. The healthcare sector has faced the need to handle the large data from different sources, renowned for generating large amounts of heterogeneous data. We can use the Big Data analysis to make proper decision in the health system by tweaking some of the current machine learning algorithms. If we have a large amount of knowledge that we want to predict or identify patterns, master learning would be the way forward. In this article, a brief overview of the Big Data, functionality and ways of Big data analytics are presented, which play an important role and affect healthcare information technology significantly. Within this paper we have presented a comparative study of algorithms for machine learning. We need to make effective use of all the current machine learning algorithms to anticipate accurate outcomes in the world of nursing.

Abstract:There is a need for some techniques to solve various problems in today's computing world. Metaheuristic algorithms are one of the techniques which are capable of providing practical solutions to such issues. Due to their efficiency, metaheuristic algorithms are now used in healthcare data to diagnose diseases practically and with better results than traditional methods. In this study, an efficient search has been performed where 173 papers from different research databases such as Scopus, Web of Science, PubMed, PsycINFO, and others have been considered impactful in diagnosing the diseases using metaheuristic techniques. Ten metaheuristic techniques have been studied, which include spider monkey, shuffled frog leaping algorithm, cuckoo search algorithm, ant lion technique of optimization, lion optimization technique, moth flame technique, bat-inspired algorithm, grey wolf algorithm, whale optimization, and dragonfly technique of optimization for selecting and optimizing the features to predict heart disease, Alzheimer's disease, brain disorder, diabetes, chronic disease features, liver disease, covid-19, etc. Besides, the framework has also been shown to provide information on various phases behind the execution of metaheuristic techniques to predict diseases. The study's primary goal is to present the contribution of the researchers by demonstrating their methodology to predict diseases using the metaheuristic techniques mentioned above. Later, their work has also been compared and evaluated using accuracy, precision, F1 score, error rate, sensitivity, specificity, an area under a curve, etc., to help the researchers to choose the right field and methods for predicting the diseases in the future.

Abstract:One of the popular metaheuristic search algorithms is Harmony Search (HS). It has been verified that HS can find solutions to optimization problems due to its balanced exploratory and convergence behavior and its simple and flexible structure. This capability makes the algorithm preferable to be applied in several real-world applications in various fields, including healthcare systems, different engineering fields, and computer science. The popularity of HS urges us to provide a comprehensive survey of the literature on HS and its variants on health systems, analyze its strengths and weaknesses, and suggest future research directions. In this review paper, the current studies and uses of harmony search are studied in four main domains. (i) The variants of HS, including its modifications and hybridization. (ii) Summary of the previous review works. (iii) Applications of HS in healthcare systems. (iv) And finally, an operational framework is proposed for the applications of HS in healthcare systems. The main contribution of this review is intended to provide a thorough examination of HS in healthcare systems while also serving as a valuable resource for prospective scholars who want to investigate or implement this method.

Abstract:The quality of service in healthcare is constantly challenged by outlier events such as pandemics (i.e. Covid-19) and natural disasters (such as hurricanes and earthquakes). In most cases, such events lead to critical uncertainties in decision making, as well as in multiple medical and economic aspects at a hospital. External (geographic) or internal factors (medical and managerial), lead to shifts in planning and budgeting, but most importantly, reduces confidence in conventional processes. In some cases, support from other hospitals proves necessary, which exacerbates the planning aspect. This manuscript presents three data-driven methods that provide data-driven indicators to help healthcare managers organize their economics and identify the most optimum plan for resources allocation and sharing. Conventional decision-making methods fall short in recommending validated policies for managers. Using reinforcement learning, genetic algorithms, traveling salesman, and clustering, we experimented with different healthcare variables and presented tools and outcomes that could be applied at health institutes. Experiments are performed; the results are recorded, evaluated, and presented.
A Survey on Optimization and Machine Learning-Based Fair Decision Making in Healthcare

Abstract:The unintended biases introduced by optimization and machine learning (ML) models are a topic of great interest to medical professionals. Bias in healthcare decisions can cause patients from vulnerable populations (e.g., racially minoritized, low-income, or living in rural areas) to have lower access to resources and inferior outcomes, thus exacerbating societal unfairness. In this systematic literature review, we present a structured overview of the literature regarding fair decision making in healthcare until April 2024. After screening 782 unique references, we identified 103 articles within the scope of our review. We categorize the identified articles into the following three sections: algorithmic bias, fairness metrics, and bias mitigation techniques. Specifically, we identify examples of algorithmic, data, and publication bias as they are typically encountered in research and practice. Subsequently, we define and discuss the fairness metrics previously considered in the literature, including notions of fairness through unawareness, demographic parity, equal opportunity, and equal odds. Lastly, we summarize the bias mitigation techniques available in the optimization and ML literature by classifying them into pre-processing, in-processing, and post-processing approaches. Fairness in decision making is an emerging field, poised to substantially reduce social inequities and improve the overall well-being of underrepresented groups. Our review aims to increase awareness of fairness in healthcare decision making and facilitate the selection of appropriate approaches under varying scenarios. Alternative Mathematical Formulation and Hybrid Meta-Heuristics for Patient Scheduling Problem in Health Care Clinics

Abstract:The proper management of patients’ waiting time requires the use of reasonable decision logic and tool. Simulation and optimization techniques can support management decisions to reduce the risk of the decision process by evaluating and analyzing various patient flow control strategies. The purpose of this study is to propose mathematical models and algorithmic frameworks to minimize the waiting time of patients and to determine the timing of the services of an emergency center. The patient scheduling problem is formulated as integer programming models, and the large instances of the problem are solved by Tabu search method and L-shaped algorithm. This cross-sectional descriptive study is conducted on 150 patients referred to the emergency department of a government hospital, and the required data are collected through a questionnaire. A discrete-event simulation model is also designed using the Arena software. According to the results of this paper, to reduce the waiting time of patients, execution of the triage process of patients in the emergency department, the use of an emergency medicine specialist for medical diagnosis and ordering the diagnostic procedures in the early stages of the process—as well as a specialist laboratory for emergency patients—are suggested to accelerate the hospital process. In the secondary work, we extended a first come first serve algorithm using a fairness ratio. The extended system prioritized the entry patients and separated non-urgent from others in terms of frequency. The result of the numerical experiments shows that the implementation of the system in five scenarios results in 11% decrement in operation time.

Abstract:Smart healthcare network is an innovative process of synergizing the benefits of sensors, Internet of things (IoT), and big data analytics to deliver improved patient care while reducing the healthcare costs. In recent days, healthcare industry faces vast challenges to save the data generated and to process it in order to extract knowledge out of it. The increasing volume of healthcare data generated through IoT devices, electronic health, mobile health, and telemedicines screening requires the development of new methods and approaches for their handling. In this chapter, we briefly discuss some of the healthcare challenges and big data analytics evolution in this fast-growing area of research with a focus on those addressed to smart health care through remote monitoring. In order to monitor the healthcare conditions of an individual, support from sensor and IoT devices is essential. The objective of this study is to provide healthcare services to the diseased as well as healthy population through remote monitoring using intelligent algorithms, tools, and techniques with faster analysis and expert intervention for better treatment recommendations. The delivery of healthcare services has become fully advanced with integration of technologies. This study proposes a novel smart healthcare big data framework for remotely monitoring physical daily activities of healthy and unhealthy population. The framework is validated through a case study which monitors the physical activities of athletes with sensors placed on wrist, chest, and ankle. The sensors connected to the human body transmit the signals continuously to the receiver. On the other hand, at the receiver end, the signals that are stored and analyzed through big data analytics techniques and machine learning algorithms are used to recognize the activity. Our proposed framework predicts whether the player is active or inactive based on the physical activities. Our proposed model has provided an accuracy of 99.96% which can be adapted to remotely monitor health conditions of old patients in case of Alzheimer’s disease by caregivers, rehabilitation, obesity monitoring, remotely monitoring of sports persons physical exertion, and it can also be beneficial for remotely monitoring chronic diseases which require vital physical information, biological, and genetic data.

Abstract:Since its inception in the early 1980s, we have seen a lot of exciting developments in the field of metaheuristics. The complexity of many real-world problems, which are often associated with large search spaces, real-time performance demands and dynamic environments, has made exact solution methods impractical to solve them within a reasonable amount of time. This gives rise to various types of non-exact metaheuristic approaches, including the natureinspired and non nature-inspired ones (see [1–4]). In general, metaheuristics can be viewed as higher level frameworks aimed at efficiently and effectively exploring a search space [5]. Unlike conventional methods, which assume that the objective functions can be solved mathematically, metaheuristics typically do not make much assumption about the problem to be solved or the underlying search space. This makes them applicable to a wide domain of tasks where little information is known about the characteristics of the utility measure. Among the most well-known metaheuristic approaches are those based on the process of natural selection, such as Genetic Algorithms (GA), Genetic Programming (GP), Evolution Strategies (ES), Evolutionary Programming (EP) and Differential Evolution (DE). Other popular metaheuristics include Simulated Annealing that takes inspiration from physics and Swarm Intelligence algorithms such as Ant Colony Optimization (ACO) and Particle Swarm Optimization (PSO) that imitate the social behavior of ants or birds. Scatter Search and Tabu Search are examples of non nature-inspired metaheuristics. These metaheuristics have been applied to areas as diverse as chemistry, computer graphics and visual arts, computer security, data mining, distributed systems, learning and teaching, economics and finance, engineering, healthcare, telecommunication networks, transportation and logistics, manufacturing, military and defense, production, and other combinatorial optimization problems. Ever since the publication of the No Free Lunch theorem [6], a theoretical result proving that the performance of every optimization algorithm over all possible (finite) problems is the same, researchers and practitioners alike have radically changed their view about designing and developing modern search heuristics. Instead of trying to propose universally applicable algorithms, they now start to propose approaches that are tailored to specific problems. Following the trend, this special issue brings together four papers in which the use of metaheuristics in specific application domains is discussed. Three of the papers included were among the invited submissions from the Special Session on Evolutionary Computing that was held at the 9th IEEE International Conference on Cognitive Informatics (ICCI 2010), Tsinghua University, Beijing, China [7]. Each of these papers was substantially revised and extended based on the original conference version. Abstract:Background: Healthcare is crucial to patient care because it provides vital services for maintaining and restoring health. As healthcare technology evolves, cutting-edge tools facilitate faster diagnosis and more effective patient treatment. In the present age of pandemics, the Internet of Things (IoT) offers a potential solution to the problem of patient safety monitoring by creating a massive quantity of data about the patient through the linked devices around them and then analyzing it to estimate the patient's current status. Utilizing the IoT-based meta-heuristic algorithm allows patients to be remotely monitored, resulting in timely diagnosis and improved care. Meta-heuristic algorithms are successful, resilient, and effective in solving real-world enhancement, clustering, predicting, and grouping. Healthcare organizations need an efficient method for dealing with big data since the prevalence of such data makes it challenging to analyze for diagnosis. The current techniques used in medical diagnostics have limitations due to imbalanced data and the overfitting issue. Objective: This study introduces the particle swarm optimization and convolutional neural network to be used as a meta-heuristic optimization method for extensive data analysis in the IoT to monitor patients' health conditions. Method: Particle Swarm Optimization is used to optimize the data used in the study. Information for a diabetes diagnosis model that includes cardiac risk forecasting is collected. Particle Swarm Optimization and Convolutional Neural Networks (PSO-CNN) results effectively make illness predictions. Support Vector Machine has been used to predict the possibility of a heart attack based on the classification of the collected data into projected abnormal and normal ranges for diabetes. Results: The results of the simulations reveal that the PSO-CNN model used to predict diabetic disease increased in accuracy by 92.6%, precision by 92.5%, recall by 93.2%, F1-score by 94.2%, and quantization error by 4.1%. Conclusion: The suggested approach could be applied to identify cancer cells.

Abstract:Big data analytics is a rapidly expanding issue in computer engineering, and health informatics is one of the most challenging topics. Big data investigation in healthcare could certainly make improvements to medical study as well as the quality of treatment offered to patients. Machine Learning (ML) algorithms due to powerful and efficient handling of data analytics could gain knowledge from data to discover patterns and trends in the database to make predictive models. Our study aims to review the most recent scholarly publications about big data analytics and its applications which include predictive models in healthcare. A systematic search of articles in the three most significant scientific databases: ScienceDirect, PubMed, and IEEE Xplore was carried out following the PRISMA methodology. This study shows how machine learning algorithms are evolving into a promising field for supporting intelligent decisions by analyzing large data sets and thereby improving treatments while reducing costs. However, there remain challenges to overcome and there is still room for improvement to develop methods and applications. Finally, we outline the unsolved issue and the future perspectives for health sciences in the big data era.

Abstract:Optimization plays an important role in tackling public health problems. Animal instincts can be used effectively to solve complex public health management issues by providing optimal or approximately optimal solutions to complicated optimization problems common in public health. BAT algorithm is an exemplary member of a class of nature-inspired metaheuristic optimization algorithms and designed to outperform existing metaheuristic algorithms in terms of efficiency and accuracy. It's inspiration comes from the foraging behavior of group of microbats that use echolocation to find their target in the surrounding environment. In recent years, BAT algorithm has been extensively used by researchers in the area of optimization, and various variants of BAT algorithm have been developed to improve its performance and extend its application to diverse disciplines. This paper first reviews the basic BAT algorithm and its variants, including their applications in various fields. As a specific application, we apply the BAT algorithm to a biostatistical estimation problem and show it has some clear advantages over existing algorithms.

Abstract:Patient triage at emergency departments (EDs) is necessary to prioritize care for patients with critical and time-sensitive conditions. In this paper, the metaheuristic optimization algorithms simulated annealing (SA) and adaptive simulated annealing (ASA) are proposed to optimize the parameters of extreme gradient boosting (XGB) and categorical boosting (CaB). The proposed algorithms are SA-XGB, ASA-XGB, SA-CaB, and ASA-CaB. Grid search (GS), a traditional approach used for machine learning fine-tuning, is also used to fine-tune the parameters of XGB and CaB, which are named GS-XGB and GS-CaB. The optimized model is used to develop an e-triage tool that can be used at EDs to predict ED patients' emergency severity index (ESI). The results show ASA-CaB outperformed all the proposed algorithms with accuracy, precision, recall, and f1 of 83.3%, 83.2%, 83.3%, and 83.2%, respectively.

Abstract:Nature-inspired metaheuristic algorithms are important components of artificial intelligence, and are increasingly used across disciplines to tackle various types of challenging optimization problems. This paper demonstrates the usefulness of such algorithms for solving a variety of challenging optimization problems in statistics using a nature-inspired metaheuristic algorithm called competitive swarm optimizer with mutated agents (CSO-MA). This algorithm was proposed by one of the authors and its superior performance relative to many of its competitors had been demonstrated in earlier work and again in this paper. The main goal of this paper is to show a typical nature-inspired metaheuristic algorithmi, like CSO-MA, is efficient for tackling many different types of optimization problems in statistics. Our applications are new and include finding maximum likelihood estimates of parameters in a single cell generalized trend model to study pseudotime in bioinformatics, estimating parameters in the commonly used Rasch model in education research, finding M-estimates for a Cox regression in a Markov renewal model, performing matrix completion tasks to impute missing data for a two compartment model, and selecting variables optimally in an ecology problem in China. To further demonstrate the flexibility of metaheuristics, we also find an optimal design for a car refueling experiment in the auto industry using a logistic model with multiple interacting factors. In addition, we show that metaheuristics can sometimes outperform optimization algorithms commonly used in statistics.

Abstract:The outbreak of chronic diseases such as COVID-19 has made a renewed call for providing urgent healthcare facilities to the citizens across the globe. The recent pandemic exposes the shortcomings of traditional healthcare system, i.e., hospitals and clinics alone are not capable to cope with this situation. One of the major technology that aids contemporary healthcare solutions is the smart and connected wearables. The advancement in Internet of Things (IoT) has enabled these wearables to collect data on an unprecedented scale. These wearables gather context-oriented information related to our physical, behavioural and psychological health. The big data generated by wearables and other healthcare devices of IoT is a challenging task to manage that can negatively affect the inference process at the decision centres. Applying big data analytics for mining information, extracting knowledge and making predictions/inferences has recently attracted significant attention. Machine learning is another area of research that has successfully been applied to solve various networking problems such as routing, traffic engineering, resource allocation, and security. Recently, we have seen a surge in the application of ML-based techniques for the improvement of various IoT applications. Although, big data analytics and machine learning are extensively researched, there is a lack of study that exclusively focus on the evolution of ML-based techniques for big data analysis in the IoT healthcare sector. In this paper, we have presented a comprehensive review on the application of machine learning techniques for big data analysis in the healthcare sector. Furthermore, strength and weaknesses of existing techniques along with various research challenges are highlighted. Our study will provide an insight for healthcare practitioners and government agencies to keep themselves well-equipped with the latest trends in ML-based big data analytics for smart healthcare.
