Abstract:This paper proposes a novel framework of writer adaptation based on deeply learned features for online handwritten Chinese character recognition. Our motivation is to further boost the state-of-the-art deep learning-based recognizer by using writer adaptation techniques. First, to perform an effective and flexible writer adaptation, we propose a tandem architecture design for the feature extraction and classification. Specifically, a deep neural network (DNN) or convolutional neural network (CNN) is adopted to extract the deeply learned features which are used to build a discriminatively trained prototype-based classifier initialized by Linde–Buzo–Gray clustering techniques. In this way, the feature extractor can fully utilize the useful information of a DNN or CNN. Meanwhile, the prototype-based classifier could be designed more compact and efficient as a practical solution. Second, the writer adaption is performed via a linear transformation of the deeply learned features which is optimized with a sample separation margin-based minimum classification error criterion. Furthermore, we improve the generalization capability of the previously proposed discriminative linear regression approach for writer adaptation by using the linear interpolation of two transformations and adaptation data perturbation. The experiments on the tasks of both the CASIA-OLHWDB benchmark and an in-house corpus with a vocabulary of 20,936 characters demonstrate the effectiveness of our proposed approach.

Abstract:This paper presents a novel approach to writer adaptation using bottleneck features and discriminative linear regression for the recognition of online handwritten Chinese characters. First, bottleneck features extracted from a bottleneck layer of a deep neural network representing a nonlinear and discriminative transformation of the input features are verified to be much more effective in adaptation of writing styles than the conventional features after linear discriminant analysis transformation. Second, discriminative linear regression via a so-called sample separation margin based minimum classification error criterion is adopted for writer adaptation. The experiments on an in-house developed online Chinese handwriting corpus with a vocabulary of 15,167 characters and testing data collected from user inputs of Smartphones show that our proposed approach can achieve very significant improvements of recognition accuracy compared with a state-of-the-art adaptation approach for writer adaptation.

Abstract:This paper presents a novel approach to writer adaptation based on convolutional neural network (CNN) as a feature extractor and improved discriminative linear regression for online handwritten Chinese character recognition. First, the proposed recognizer consisting of CNN-based feature extractor and prototype-based classifier can achieve comparable performance with the state-of-the-art CNN-based classifier while it could be designed more compact and efficient as a practical solution. Second, the writer adaption is performed via a linear transformation of the extracted feature from CNN. The transformation parameters are optimized with a so-called sample separation margin based minimum classification error criterion, which can be further improved by using more synthesized adaptation data and a simple regularization method. The experiments on the data collected from user inputs of Smartphones with a vocabulary of 20,936 characters demonstrate that our writer adaptation approach can yield significant improvements of recognition accuracy over a high-performance baseline system and also outperform a state-of-the-art approach based on style transfer mapping especially with increased adaptation data.
Off- Line Chinese Writer Identification Based on Character-Level Decision Combination

Abstract:In this paper, a novel method to accelerate off-line Chinese writer identification by combining multi text-sensitive features and combining multi character level decisions is practiced. The used text-sensitive writer identification algorithm extracts Directional histogram feature, Moment feature and Wigner feature, reduces the dimensions using PCA and LDA, and adopts the simple Euclidean classifier. However the writer identification algorithms are text-sensitive, thus there are different mutual character combinations between writers. A method for retrieving in an amount of writers who has different handwriting script content is proposed in this paper, by combining and sorting the posterior probability measures of writing identification. An experiment, which is carried out in a handwriting script database, demonstrates the effectiveness of the proposed method.

Abstract:Most existing systems use portable devices or image processing techniques for handwritten Chinese character recognition (HCCR), which are unable to detect character when writing on a paper or sensitive to lighting conditions. In this article, we present the design, implementation, and evaluation of a smartwatch-based HCCR system, called SmartHandwriting. To segment each Chinese character, we further analyze the hand movement between the handwriting gesture and the wrist movement gesture and propose a novel algorithm to distinguish the two types of gestures. Due to too many Chinese characters for classification, we utilize the data augmentation method for avoiding overfitting. Then, we build the HCCR model using the deep convolutional neural network (DCNN) method. The recognition accuracy of the Chinese characters is 96.0%, and extensive experiments confirm its effectiveness and robustness. Moreover, we also explore adverse factors that affect the recognition performance, which can be avoided in the future.
Writer Code Based Adaptation of Deep Neural Network for Offline Handwritten Chinese Text Recognition.

Abstract:Recently, we propose deep neural network based hidden Markov models (DNN-HMMs)for offline handwritten Chinese text recognition. In this study, we design a novel writer code based adaptation on top of the DNN-HMM to further improve the accuracy via a customized recognizer. The writer adaptation is implemented by incorporating the new layers with the original input or hidden layers of the writer-independent DNN. These new layers are driven by the so-called writer code, which guides and adapts the DNN-based recognizer with the writer information. In the training stage, the writer-aware layers are jointly learned with the conventional DNN layers in an alternative manner. In the recognition stage, with the initial recognition results from the first-pass decoding with the writer-independent DNN, an unsupervised adaptation is performed to generate the writer code via the cross-entropy criterion for the subsequent. second-pass decoding. The experiments on the most challenging task of ICDAR 2013 Chinese handwriting competition show that our proposed adaptation approach can achieve consistent and significant improvements of recognition accuracy over a high-performance writer-independent DNN-HMM based recognizer across all 60 writers, yielding a relative character error rate reduction of 23.62% in average.

Abstract:Writing style is an abstract attribute in handwritten text. It plays an important role in recognition systems and is not easy to define explicitly. Considering the effect of writing style, a writer adaptation method is proposed to transform a writer-independent recognizer toward a particular writer. This transformation has the potential to significantly increase accuracy. In this paper, under the deep learning framework, we propose a general fast writer adaptation solution. Specifically, without depending on other complex skills, a well designed style extractor network (SEN) trained by identification loss (IDL) is introduced to explicitly extract personalized writer information. The architecture of SEN consists of a stack of convolutional layers followed by a recurrent neural network with gated recurrent units to remove semantic context and retain writer information. Then, the outputs of the GRU are further integrated into a one-dimensional vector that is adopted to represent writing style. Finally, the extracted style information is fed into the writer-independent recognizer to achieve adaptation. Validated on offline handwritten text recognition tasks, the proposed fast sentence-level adaptation achieves remarkable improvements in Chinese and English text recognition tasks. Specifically, in the HETR task, a multi-information fusion network that is equipped with a hybrid attention mechanism and that integrates visual features, context features and writing style is proposed. In addition, under the same condition (only one writer-specific text line used as adaptation data), the proposed solution, without consuming extra time, can significantly outperform the previous multiple-pass decoding method. Character-level Chinese Writer Identification using Path Signature Feature, DropStroke and Deep CNN

Abstract:Most existing online writer-identification systems require that the text content is supplied in advance and rely on separately designed features and classifiers. The identifications are based on lines of text, entire paragraphs, or entire documents; however, these materials are not always available. In this paper, we introduce a path-signature feature to an end-to-end text-independent writer-identification system with a deep convolutional neural network (DCNN). Because deep models require a considerable amount of data to achieve good performance, we propose a data-augmentation method named DropStroke to enrich personal handwriting. Experiments were conducted on online handwritten Chinese characters from the CASIA-OLHWDB1.0 dataset, which consists of 3,866 classes from 420 writers. For each writer, we only used 200 samples for training and the remaining 3,666. The results reveal that the path-signature feature is useful for writer identification, and the proposed DropStroke technique enhances the generalization and significantly improves performance.

Bag of Features Approach for Offline Text-Independent Chinese Writer Identification

Abstract:This paper studies offline text-independent writer identification of Chinese handwriting. The Bag of Features method is adopted for Chinese writer identification and performs much better than previous state-of-the-art methods. The feature adopted is scale invariant transform feature (SIFT) descriptor for it can extract local directional information from Chinese characters. Instead of Hard Voting, we use two newly devised coding strategies: Improved Fisher Kernels and Locality-constrained Linear Coding, to encode each SIFT descriptor. To make these coding strategies suitable to this new application area, absolute average pooling function is utilized. At last the K-nearest-neighbor classifier is used to identify the author of a handwriting image. Experimental results are conducted on a newly collected dataset of Chinese handwriting, CASIA Offline DB 2.1. Experimental results show our approach not only outperforms previous state-of-the-art methods, but also the traditional Bag of Word method using Hard Voting.
A Stroke-Based RNN for Writer-Independent Online Signature Verification.

Abstract:In the field of online handwritten signature verification, it is challenging to verify handwritten signature in a writer-independent scenario. In recent years, many researchers have been applying deep neural network methods to the signature verification task. However, these methods have not outperformed traditional methods, especially when the training samples are limited. In this paper, we propose a novel stroke-based bidirectional RNN architecture. The main idea is to split the signature into multiple patches using strokes. Concatenation of query and reference signature pairs are used as input. The proposed method uses two LSTM RNN networks to extract different features. The first one extracts the features of the strokes and the latter extracts the global features of the whole signatures. The results on the BiosecureID dataset demonstrate that our proposed method can reduce the EER by 33.05%, from 5.6% to 3.75% with fewer features and less training samples. Besides, we find that the proposed stroke based RNN network is 5x faster in training and testing time than Non stroke-based RNN network.

Abstract:The recurrent neural network (RNN) is appropriate for dealing with temporal sequences. In this paper, we present a deep RNN with new features and apply it for online handwritten Chinese character recognition. Compared with the existing RNN models, three innovations are involved in the proposed system. First, a new hidden layer function for RNN is proposed for learning temporal information better. we call it Memory Pool Unit (MPU). The proposed MPU has a simple architecture. Second, a new RNN architecture with hybrid parameter is presented, in order to increasing the expression capacity of RNN. The proposed hybrid-parameter RNN has parameter changes when calculating the iteration at temporal dimension. Third, we make a adaptation that all the outputs of each layer are stacked as the output of network. Stacked hidden layer states combine all the hidden layer states for increasing the expression capacity. Experiments are carried out on the IAHCC-UCAS2016 dataset and the CASIA-OLHWDB1.1 dataset. The experimental results show that the hybrid-parameter RNN obtain a better recognition performance with higher efficiency (fewer parameters and faster speed). And the proposed Memory Pool Unit is proved to be a simple hidden layer function and obtains a competitive recognition results.

Abstract:Recently Optical character recognition (OCR) based on deep learning technology has achieved great advance and broadly applied in various industries. However it still faces many challenging problems in handwritten text recognition and mathematical expression recognition, such as handwritten Chinese recognition, mixture of printed and handwritten Chinese characters, mathematical expression (ME), chemical equations. In traditional OCR, features selection played a vital role for recognition accuracy, while hand-crafted features are costly and time-consuming. In this paper, we introduce a deep learning based framework to detect and recognize handwritten and printed text or math expression. The framework consists of three components. The first component is DCN (Detection & Classification Network), which based on SSD model to detects and classify mathematical expression and text. The second component consists of text recognition and ME recognition models. The final component merges multiple outputs of the second stage into a whole text. Experiment results show that our framework achieves a relative 10% improvement in mixture of texts and MEs which are printed or handwritten in images. The framework has been deployed for recognition paper or homework at one online education platform.
Online Chinese Handwriting Recognition with Time Sequence Information

Abstract:Handwriting recognition has been a heated topic over years. Due to the development of deep learning, a lot of research has been done to apply convolutional neural network (CNN) model to this task, which have achieved outstanding accuracy. Instead of focusing merely on CNN models, this article takes the features of Chinese handwritten character into consideration and manages to extract the information of the stroke order of the online handwriting recognition. To achieve this, two methods are proposed: (1) Design a two-branch model combining CNN and recurrent neural network (RNN);(2) Give a new channel division strategy. Also, the task of advanced prediction of the character which little research has been worked on is the key point. With the information of stroke order and some data augmentation strategy, methods proposed have achieved satisfying results.
A Study of Designing Compact Classifiers Using Deep Neural Networks for Online Handwritten Chinese Character Recognition

Two schemes are investigated based on practical considerations. First, deep neural networks are adopted purely as a classifier with a state-of-the-art feature extractor of online handwritten Chinese characters. Second, the so-called bottleneck features extracted from a bottleneck layer of deep neural networks are fed to the prototype-based classifier. The experiments on an in-house developed online Chinese handwriting corpus with a vocabulary of 15,167 characters show that compared with prototype-based classifier widely developed on the mobile device, deep neural network based classifier can yield significant improvements of recognition accuracy with acceptably increased footprint and latency while the bottleneck-feature approach can bring a more compact classifier with an observable performance gain.

Abstract:Chinese characters are complex and contain discriminative information, meaning that their writers have the potential to be recognized using less text. In this study, offline Chinese writer identification based on a single character was investigated. To extract comprehensive features to model Chinese characters, explicit and implicit information as well as global and local features are of interest. A dual-branch multitask fusion network is proposed that contains two branches for global and local feature extraction simultaneously, and introduces auxiliary tasks to help the main task. Content recognition, stroke number estimation, and stroke recognition are considered as three auxiliary tasks for explicit information. The main task extracts implicit information of writer identity. The experimental results validated the positive influences of auxiliary tasks on the writer identification task, with the stroke number estimation task being most helpful. In-depth research was conducted to investigate the influencing factors in Chinese writer identification, with respect to character complexity, stroke importance, and character number, which provides a systematic reference for the actual application of neural networks in Chinese writer identification.

Abstract:Empowering machines to own the capability of writing texts as human beings has been a long-standing goal in the community. The task is challenging due to the complexity of human handwriting behaviors when writing long text lines or articles, especially for some writing systems (e.g., Chinese) that contain vast amounts of glyphs with complicated geometric appearances and structures. In this paper, we propose a novel system, CHWMaster, to mimic the behavior of an arbitrary user to write Chinese articles in the user’s personalized handwriting style. The key idea of our proposed method is to design a new model based on deep Recurrent Neural Networks with sliding windows. Both qualitative and quantitative experiments have been conducted to demonstrate that with the help of our proposed CHWMaster, for the first time, robots are able to write Chinese articles like humans, getting high-fidelity Chinese handwritten texts that are indistinguishable from real ones by simply feeding one/a few human-written text lines to fine-tune our pre-trained model.
Writer-Aware CNN for Parsimonious HMM-Based Offline Handwritten Chinese Text Recognition

Abstract:Recently, the hybrid convolutional neural network hidden Markov model (CNN-HMM) has been introduced for offline handwritten Chinese text recognition (HCTR) and has achieved state-of-the-art performance. However, modeling each of the large vocabulary of Chinese characters with a uniform and fixed number of hidden states requires high memory and computational costs and makes the tens of thousands of HMM state classes confusing. Another key issue of CNN-HMM for HCTR is the diversified writing style, which leads to model strain and a significant performance decline for specific writers. To address these issues, we propose a writer-aware CNN based on parsimonious HMM (WCNN-PHMM). First, PHMM is designed using a data-driven state-tying algorithm to greatly reduce the total number of HMM states, which not only yields a compact CNN by state sharing of the same or similar radicals among different Chinese characters but also improves the recognition accuracy due to the more accurate modeling of tied states and the lower confusion among them. Second, WCNN integrates each convolutional layer with one adaptive layer fed by a writer-dependent vector, namely, the writer code, to extract the irrelevant variability in writer information to improve recognition performance. The parameters of writer-adaptive layers are jointly optimized with other network parameters in the training stage, while a multiple-pass decoding strategy is adopted to learn the writer code and generate recognition results. Validated on the ICDAR 2013 competition of CASIA-HWDB database, the more compact WCNN-PHMM of a 7360-class vocabulary can achieve a relative character error rate (CER) reduction of 16.6% over the conventional CNN-HMM without considering language modeling. By adopting a powerful hybrid language model (N-gram language model and recurrent neural network language model), the CER of WCNN-PHMM is reduced to 3.17%.

Improved Deep Convolutional Neural Network For Online Handwritten Chinese Character Recognition using Domain-Specific Knowledge

Abstract:Deep convolutional neural networks (DCNNs) have achieved great success in various computer vision and pattern recognition applications, including those for handwritten Chinese character recognition (HCCR). However, most current DCNN-based HCCR approaches treat the handwritten sample simply as an image bitmap, ignoring some vital domain-specific information that may be useful but that cannot be learnt by traditional networks. In this paper, we propose an enhancement of the DCNN approach to online HCCR by incorporating a variety of domain-specific knowledge, including deformation, non-linear normalization, imaginary strokes, path signature, and 8-directional features. Our contribution is twofold. First, these domain-specific technologies are investigated and integrated with a DCNN to form a composite network to achieve improved performance. Second, the resulting DCNNs with diversity in their domain knowledge are combined using a hybrid serial-parallel (HSP) strategy. Consequently, we achieve a promising accuracy of 97.20% and 96.87% on CASIA-OLHWDB1.0 and CASIA-OLHWDB1.1, respectively, outperforming the best results previously reported in the literature.

Abstract:Off-screen handwriting recognition enriches the handwriting interaction paradigm for mobile devices. However, the existing approaches are only applicable to the specific environment and equipment conditions. In this paper, we propose AcouWrite, a general, scalable and real-time handwriting recognition system based on active acoustic sensing. In detail, AcouWrite relies on active acoustic sensing using only a pair of microphones and speakers on the smartphone to capture real-time handwriting input. Particularly, we extract the short-time dCIR (st-dCIR) to monitor the changes in the acoustic transmission channel resulting from finger movement. Technically, we use a CNN-GRU classifier to complete the recognition task in AcouWrite. Moreover, we use data augmentation and spelling error correction methods to improve AcouWrite's robustness. To improve the generalization of our AcouWrite for new characters, we incorporate the transfer learning module into our AcouWrite. In various real-world environments, experiments demonstrate that AcouWrite achieves a mean recognition accuracy of 97.62%, a word accuracy (WA) of 96.4% and a character error rate (CER) of 1.5% for 100 common words, and an average response time of 94 milliseconds.
