Abstract:Recently, automatic accent recognition has been paid more and more attentions. However, there are few researches focusing on accent recognition in distant-talking environment which is very important for improving distant-talking speech recognition performance with non-native accents. In this paper, we apply Gaussian Mixture Models (GMM) and Deep Neural Network (DNN) to identify the speaker accent in reverberant environments. The combination of likelihood with these two approaches is also proposed. In reverberant environment, the accent recognition rate was improved from 90.7 % with GMM to 93.0 % with DNN. The combination of GMM and DNN achieved recognition rate of 97.5 %, which outperformed than the individual GMM and DNN because the complementation of GMM and DNN. The relative error reduction is 73.1 % than the GMM-based method and 64.3 % than the DNN-based method, respectively.
Multilingual Approach to Joint Speech and Accent Recognition with DNN-HMM Framework

Abstract:Human can recognize speech, as well as the peculiar accent of the speech simultaneously. However, present state-of-the-art ASR system can rarely do that. In this paper, we propose a multilingual approach to recognizing English speech, and related accent that speaker conveys using DNN-HMM framework. Specifically, we assume different accents of English as different languages. We then merge them together and train a multilingual ASR system. During decoding, we conduct two experiments. One is a monolingual ASR-based decoding, with the accent information embedded at phone level, realizing word-based accent recognition (AR), and the other is a multilingual ASR-based decoding, realizing an approximated utterance-based AR. Experimental results on an 8-accent English speech recognition show both methods can yield WERs close to the conventional ASR systems that completely ignore the accent, as well as desired AR accuracy. Besides, we conduct extensive analysis for the proposed method, such as transfer learning without-domain data exploitation, cross-accent recognition confusion, as well as characteristics of accented-word.

Deep Neural Network-Based Bottleneck Feature and Denoising Autoencoder-Based Dereverberation for Distant-Talking Speaker Identification.

Abstract:Deep neural network (DNN)-based approaches have been shown to be effective in many automatic speech recognition systems. However, few works have focused on DNNs for distant-talking speaker recognition. In this study, a bottleneck feature derived from a DNN and a cepstral domain denoising autoencoder (DAE)-based dereverberation are presented for distant-talking speaker identification, and a combination of these two approaches is proposed. For the DNN-based bottleneck feature, we noted that DNNs can transform the reverberant speech feature to a new feature space with greater discriminative classification ability for distant-talking speaker recognition. Conversely, cepstral domain DAE-based dereverberation tries to suppress the reverberation by mapping the cepstrum of reverberant speech to that of clean speech with the expectation of improving the performance of distant-talking speaker recognition. Since the DNN-based discriminant bottleneck feature and DAE-based dereverberation have a strong complementary nature, the combination of these two methods is expected to be very effective for distant-talking speaker identification. A speaker identification experiment was performed on a distant-talking speech set, with reverberant environments differing from the training environments. In suppressing late reverberation, our method outperformed some state-of-the-art dereverberation approaches such as the multichannel least mean squares (MCLMS). Compared with the MCLMS, we obtained a reduction in relative error rates of 21.4% for the bottleneck feature and 47.0% for the autoencoder feature. Moreover, the combination of likelihoods of the DNN-based bottleneck feature and DAE-based dereverberation further improved the performance.
Emphasis Detection for Voice Dialogue Applications Using Multi-channel Convolutional Bidirectional Long Short-Term Memory Network

Abstract:Emphasis detection is important for user intention understanding in human-computer interaction scenario. Techniques have been developed to detect the emphatic words in speech, but challenges still exist in Voice Dialogue Applications (VDAs): the tremendous non-specific speakers and their various expressions. In this work, we present a novel approach to automatically detect emphasis in VDAs by using multi-channel convolutional bi -directional long short-term memory neural networks (MC-BLSTM), which can learn various expressions of large amounts of speakers and long span temporal dependencies across speech trajectories. In particular, we first use a multi-channel convolutional component in the proposed approach to extract high-level representation of input acoustic features for emphasis detection. The experimental results on a 3400 real-world dataset collected from Sogou 11http://yy.sogou.com Voice Assistant outper-form current state-of-the-art baseline systems (+6.2% in terms of F1-measure on average).
Phonotactic language recognition based on DNN-HMM acoustic model

Abstract:A recently introduced deep neural network (DNN) has achieved some unprecedented gains in many challenging automatic speech recognition (ASR) tasks. In this paper deep neural network hidden Markov model (DNN-HMM) acoustic models is introduced to phonotactic language recognition and outperforms artificial neural network hidden Markov model (ANN-HMM) and Gaussian mixture model hidden Markov model (GMM-HMM) acoustic model. Experimental results have confirmed that phonotactic language recognition system using DNN-HMM acoustic model yields relative equal error rate reduction of 28.42%, 14.06%, 18.70% and 12.55%, 7.20%, 2.47% for 30s, 10s, 3s comparing with the ANN-HMM and GMM-HMM approaches respectively on National Institute of Standards and Technology language recognition evaluation (NIST LRE) 2009 tasks.
Inferring Emphasis for Real Voice Data: an Attentive Multimodal Neural Network Approach.

Abstract:To understand speakers’ attitudes and intentions in real Voice Dialogue Applications (VDAs), effective emphasis inference from users’ queries may play an important role. However, in VDAs, there are tremendous amount of uncertain speakers with a great diversity of users’ dialects, expression preferences, which challenge the traditional emphasis detection methods. In this paper, to better infer emphasis for real voice data, we propose an attentive multimodal neural network. Specifically, first, beside the acoustic features, extensive textual features are applied in modelling. Then, considering the feature in-dependency, we model the multi-modal features utilizing a Multi-path convolutional neural network (MCNN). Furthermore, combining high-level multi-modal features, we train an emphasis classifier by attending on the textual features with an attention-based bidirectional long short-term memory network (ABLSTM), to comprehensively learn discriminative features from diverse users. Our experimental study based on a real-world dataset collected from Sogou Voice Assistant ( https://yy.sogou.com/ ) show that our method outperforms (over 1.0–15.5% in terms of F1 measure) alternative baselines.

Abstract:State-of-the-art automatic speech recognition models often struggle to capture nuanced features inherent in accented speech, leading to sub-optimal performance in speaker recognition based on regional accents. Despite substantial progress in the field of automatic speech recognition, ensuring robustness to accents and generalization across dialects remains a persistent challenge, particularly in real-time settings. In response, this study introduces a novel approach leveraging Variational Mode Decomposition (VMD) to enhance accented speech signals, aiming to mitigate noise interference and improve generalization on unseen accented speech datasets. Our method employs decomposed modes of the VMD algorithm for signal reconstruction, followed by feature extraction using Mel-Frequency Cepstral Coefficients (MFCC). These features are subsequently classified using machine learning models such as 1D Convolutional Neural Network (1D-CNN), Support Vector Machine (SVM), Random Forest, and Decision Trees, as well as a deep learning model based on a 2D Convolutional Neural Network (2D-CNN). Experimental results demonstrate superior performance, with the SVM classifier achieving an accuracy of approximately 87.5% on a standard dataset and 99.3% on the AccentBase dataset. The 2D-CNN model further improves the results in multi-class accent classification tasks. This research contributes to advancing automatic speech recognition robustness and accent-inclusive speaker recognition, addressing critical challenges in real-world applications.

Deep Discriminative Feature Learning for Accent Recognition

Abstract:Accent recognition with deep learning framework is a similar work to deep speaker identification, they’re both expected to give the input speech an identifiable representation. Compared with the individual-level features learned by speaker identification network, the deep accent recognition work throws a more challenging point that forging group-level accent features for speakers. In this paper, we borrow and improve the deep speaker identification framework to recognize accents, in detail, we adopt Convolutional Recurrent Neural Network as frontend encoder and integrate local features using Recurrent Neural Network to make an utterance-level accent representation. Novelly, to address overfitting, we simply add Connectionist Temporal Classification based speech recognition auxiliary task during training, and for ambiguous accent discrimination, we introduce some powerful discriminative loss functions in face recognition works to enhance the discriminative power of accent features. We show that our proposed network with discriminative training method (without data-augment) is significantly ahead of the baseline system on the accent classification track in the Accented English Speech Recognition Challenge 2020, where the loss function Circle-Loss has achieved the best discriminative optimization for accent representation.
Improved Accent Classification Combining Phonetic Vowels with Acoustic Features

Abstract:Researches have shown accent classification can be improved by integrating semantic information into pure acoustic approach. In this work, we combine phonetic knowledge, such as vowels, with enhanced acoustic features to build an improved accent classification system. The classifier is based on Gaussian Mixture Model-Universal Background Model (GMM-UBM), with normalized Perceptual Linear Predictive (PLP) features. The features are further optimized by Principle Component Analysis (PCA) and Hetroscedastic Linear Discriminant Analysis (HLDA). Using 7 major types of accented speech from the Foreign Accented English (FAE) corpus, the system achieves classification accuracy 54% with input test data as short as 20 seconds, which is competitive to the state of the art in this field.
A Study of Enhancement, Augmentation, and Autoencoder Methods for Domain Adaptation in Distant Speech Recognition

Abstract:Speech recognizers trained on close-talking speech do not generalize to distant speech and the word error rate degradation can be as large as 40% absolute. Most studies focus on tackling distant speech recognition as a separate problem, leaving little effort to adapting close-talking speech recognizers to distant speech. In this work, we review several approaches from a domain adaptation perspective. These approaches, including speech enhancement, multi-condition training, data augmentation, and autoencoders, all involve a transformation of the data between domains. We conduct experiments on the AMI data set, where these approaches can be realized under the same controlled setting. These approaches lead to different amounts of improvement under their respective assumptions. The purpose of this paper is to quantify and characterize the performance gap between the two domains, setting up the basis for studying adaptation of speech recognizers from close-talking speech to distant speech. Our results also have implications for improving distant speech recognition.

Speech Selection and Environmental Adaptation for Asynchronous Speech Recognition

Abstract:In this paper, we propose a robust distant-talking speech recognition system with asynchronous speech recording. This is implemented by combining automatic asynchronous speech (microphone or mobile terminal) selection and environmental adaptation with deep neural network based framework. Although applications using mobile terminals have attracted increasing attention, there are few studies that focus on distant-talking speech recognition with asynchronous mobile terminals. For the system proposed in this paper, by using bottleneck Features (BFs) from a Deep Neural Network (DNN) rather than the conventional Mel-Frequency Cesptral Coefficients (MFCCs), we adopted the state-of-the-art deep neural network acoustic model, environmental adaptation and automatic asynchronous speech selection. The proposed method was evaluated by using a reverberant WSJCAM0 corpus, which was emitted by a loudspeaker and recorded in a meeting room with multiple speakers by far-field multiple mobile terminals. By using the bottleneck features based DNN acoustic model with automatic asynchronous speech selection and environmental adaptation, the average Word Error Rate (WER) was reduced from 55.32% of the baseline system to 19.38%, i.e. the relative error reduction rate was 64.97%.
Mandarin accent identification based on GMM with multi-feature fusion

Abstract:A method based on Mel frequency cepstrum coefficients (MFCC) and formant frequency for Mandarin accent identification was proposed. Firstly, MFCC and formant frequency features were extracted for the Gaussian mixture model (GMM), which was trained by the expectation-maximization (EM) algorithm. Then, these two features were modeled. Finally, the information fusion strategy based on maximum likelihood (ML) criteria was utilized to make the final decision. The corpus consists of speech data from seven districts. After cross-validation, the results indicate that the recognition rate can reach 85.61% for the typical parts of Mandarin-speaking areas in China. Compared with the approaches of using MFCC or formant frequency features, our method increases by 6.62% and 32.90%, respectively. ©, 2015, Huazhong University of Science and Technology. Foreign English Accent Adjustment by Learning Phonetic Patterns

Abstract:State-of-the-art automatic speech recognition (ASR) systems struggle with the lack of data for rare accents. For sufficiently large datasets, neural engines tend to outshine statistical models in most natural language processing problems. However, a speech accent remains a challenge for both approaches. Phonologists manually create general rules describing a speaker's accent, but their results remain underutilized. In this paper, we propose a model that automatically retrieves phonological generalizations from a small dataset. This method leverages the difference in pronunciation between a particular dialect and General American English (GAE) and creates new accented samples of words. The proposed model is able to learn all generalizations that previously were manually obtained by phonologists. We use this statistical method to generate a million phonological variations of words from the CMU Pronouncing Dictionary and train a sequence-to-sequence RNN to recognize accented words with 59% accuracy.

Distant-talking Speaker Identification by Generalized Spectral Subtraction-Based Dereverberation and Its Efficient Computation

Abstract:Previously, a dereverberation method based on generalized spectral subtraction (GSS) using multi-channel least mean-squares (MCLMS) has been proposed. The results of speech recognition experiments showed that this method achieved a significant improvement over conventional methods. In this paper, we apply this method to distant-talking (far-field) speaker recognition. However, for far-field speech, the GSS-based dereverberation method using clean speech models degrades the speaker recognition performance. This may be because GSS-based dereverberation causes some distortion between clean speech and dereverberant speech. In this paper, we address this problem by training speaker models using dereverberant speech obtained by suppressing reverberation from arbitrary artificial reverberant speech. Furthermore, we propose an efficient computational method for a combination of the likelihood of dereverberant speech using multiple compensation parameter sets. This addresses the problem of determining optimal compensation parameters for GSS. We report the results of a speaker recognition experiment performed on large-scale far-field speech with different reverberant environments to the training environments. The proposed GSS-based dereverberation method achieves a recognition rate of 92.2%, which compares well with conventional cepstral mean normalization with delay-and-sum beamforming using a clean speech model (49.0%) and a reverberant speech model (88.4%). We also compare the proposed method with another dereverberation technique, multi-step linear prediction-based spectral subtraction (MSLP-GSS). The proposed method achieves a better recognition rate than the 90.6% of MSLP-GSS. The use of multiple compensation parameters further improves the speech recognition performance, giving our approach a recognition rate of 93.6%. We implement this method in a real environment using the optimal compensation parameters estimated from an artificial environment. The results show a recognition rate of 87.8% compared with 72.5% for delay-and-sum beamforming using a reverberant speech model.
Automatic lexical stress and pitch accent detection for L2 English speech using multi-distribution deep neural networks

Abstract:This paper investigates the use of multi-distribution deep neural networks (MD-DNNs) for automatic lexical stress detection and pitch accent detection, which are useful for suprasegmental mispronunciation detection and diagnosis in second-language (L2) English speech. The features used in this paper cover syllable-based prosodic features (including maximum syllable loudness, syllable nucleus duration and a pair of dynamic pitch values) as well as lexical and syntactic features (encoded as binary variables). As stressed/accented syllables are more prominent than their neighbors, the two preceding and two following syllables are also taken into consideration. Experimental results show that the MD-DNN for lexical stress detection achieves an accuracy of 87.9% in syllable classification (primary/secondary/no stress) for words with three or more syllables. This performance is much better than those of our previous work using Gaussian mixture models (GMMs) and the prominence model (PM), whose accuracies are 72.1% and 76.3% respectively. Approached similarly as the lexical stress detector, the pitch accent detector obtains an accuracy of 90.2%, which is better than the results of using the GMMs and PM by about 9.6% and 6.9% respectively.

Investigation of Deep Neural Network Acoustic Modelling Approaches for Low Resource Accented Mandarin Speech Recognition

Abstract:The Mandarin Chinese language is known to be strongly influenced by a rich set of regional accents, while Mandarin speech with each accent is quite low resource. Hence, an important task in Mandarin speech recognition is to appropriately model the acoustic variabilities imposed by accents. In this paper, an investigation of implicit and explicit use of accent information on a range of deep neural network (DNN) based acoustic modelling techniques is conducted. Meanwhile, approaches of multi-accent modelling including multi-style training, multi-accent decision tree state tying, DNN tandem and multi-level adaptive network (MLAN) tandem hidden Markov model (HMM) modelling are combined and compared in this paper. On a low resource accented Mandarin speech recognition task consisting of four regional accents, an improved MLAN tandem HMM systems explicitly leveraging the accent information was proposed and significantly outperformed the baseline accent independent DNN tandem systems by 0.8%-1.5% absolute (6%-9% relative) in character error rate after sequence level discriminative training and adaptation.

Reliable accent specific unit generation with dynamic Gaussian mixture selection for multi-accent speech recognition

Abstract:Multiple accents are often present in Mandarin speech, as most Chinese have learned Mandarin as a second language. We propose generating reliable accent specific unit together with dynamic Gaussian mixture selection for multi-accent speech recognition. Time alignment phoneme recognition is used to generate such unit and to model accent variations explicitly and accurately. Dynamic Gaussian mixture selection scheme builds a dynamical observation density for each specified frame in decoding, and leads to use Gaussian mixture component efficiently. This method increases the covering ability for a diversity of accent variations in multi-accent, and alleviates the performance degradation caused by pruned beam search without augmenting the model size. The effectiveness of this approach is evaluated on three typical Chinese accents Chuan, Yue and Wu. Our approach outperforms traditional acoustic model reconstruction approach significantly by 6.30%, 4.93% and 5.53%, respectively on Syllable Error Rate (SER) reduction, without degrading on standard speech.
Joint Training of DNNs by Incorporating an Explicit Dereverberation Structure for Distant Speech Recognition

Abstract:We explore joint training strategies of DNNs for simultaneous dereverberation and acoustic modeling to improve the performance of distant speech recognition. There are two key contributions. First, a new DNN structure incorporating both dereverberated and original reverberant features is shown to effectively improve recognition accuracy over the conventional one using only dereverberated features as the input. Second, in most of the simulated reverberant environments for training data collection and DNN-based dereverberation, the resource data and learning targets are high-quality clean speech. With our joint training strategy, we can relax this constraint by using large-scale diversified real close-talking data as the targets which are easy to be collected via many speech-enabled applications from mobile internet users, and find the scenario even more effective. Our experiments on a Mandarin speech recognition task with 2000-h training data show that the proposed framework achieves relative word error rate reductions of 9.7 and 8.6 % over the multi-condition training systems for the cases of single-channel and multi-channel with beamforming, respectively. Furthermore, significant gains are consistently observed over the pre-processing approach using simply DNN-based dereverberation.

Abstract:We propose an attribute-based approach to accented speech recognition based on automatic speech attribute transcription with high efficiency detection of articulatory features. In order to utilize appropriate and extensible phonetic and linguistic knowledge, conditional random field (CRF) is designed to take frame-level inputs with binary feature functions. The use of CRF with merely the state features to generate probabilistic phone lattices is then utilized to solve the phone under-generation problem. Finally an attribute discrimination module is incorporated to handle a diversity of accent changes without retraining any model, leading to flexible "plug 'n' play" modular design. The effectiveness of the proposed approach is evaluated on three typical Chinese accents, namely Guanhua, Yue and Wu. Our method yields a significant absolute phone recognition accuracy improvement 5.04%, 4.68% and 6.06% for the corresponding three accent types over a conventional monophone HMM system. Compared to a context-dependent triphone HMM system, we achieve comparable phone accuracies at only less than 20% of the computation cost. In addition, our proposed method is equally applicable to speaker-independent systems handling multiple accents. © 2011 IEEE.
