Abstract:In order to process complex and large-scale graph data numerous distributed graph-parallel computing platforms have been proposed. However, excessive communications among computing nodes in these systems not only aggravate the network I/O workload of the underlying computing hardware systems but may also cause a decrease in runtime performance and scalability. In this paper, we propose and implement a system called Ligraph, which computes large-scale graph data in distributed mode with lightweight communication overhead. Ligraph is similar to PowerGraph system with three new features: (1) a Gather partial sum difference based computing model; (2) a corresponding lightweight Gather communication mechanism; (3) for PageRank-like algorithms Ligraph additionally employs a lightweight synchronizing communication mechanism and an edge direction-aware graph partition strategy proposed by our former work LightGraph, which is specially designed for PageRank-like algorithms. We have conducted extensive experiments using real-world data sets, and our results verified the effectiveness of Ligraph on reducing the communication overhead and improving the runtime performance and the scalability compared with PowerGraph and LightGraph. For example, compared with PowerGraph under Random partition scenario Ligraph can not only reduce up to 35.2 percent of the communication overhead but also cut up to 21.8 percent of the runtime for PageRank algorithm while processing Twitter data set. Our experiment results also demonstrate that compared with several other representative existing systems Ligraph also outperforms them in graph computing rate.
DGCC: A New Dependency Graph based Concurrency Control Protocol for Multicore Database Systems.

Abstract: Multicore CPUs and large memories are increasingly becoming the norm in modern computer systems. However, current database management systems (DBMSs) are generally ineffective in exploiting the parallelism of such systems. In particular, contention can lead to a dramatic fall in performance. In this paper, we propose a new concurrency control protocol called DGCC (Dependency Graph based Concurrency Control) that separates concurrency control from execution. DGCC builds dependency graphs for batched transactions before executing them. Using these graphs, contentions within the same batch of transactions are resolved before execution. As a result, the execution of the transactions does not need to deal with contention while maintaining full equivalence to that of serialized execution. This better exploits multicore hardware and achieves higher level of parallelism. To facilitate DGCC, we have also proposed a system architecture that does not have certain centralized control components yielding better scalability, as well as supports a more efficient recovery mechanism. Our extensive experimental study shows that DGCC achieves up to four times higher throughput compared to that of state-of-the-art concurrency control protocols for high contention workloads.
Graph Analytics Through Fine-Grained Parallelism.

Abstract:Large graphs are getting increasingly popular and even indispensable in many applications, for example, in social media data, large networks, and knowledge bases. Efficient graph analytics thus becomes an important subject of study. To increase efficiency and scalability, in-memory computation and parallelism have been explored extensively to speed up various graph analytical workloads. In many graph analytical engines (e.g., Pregel, Neo4j, GraphLab), parallelism is achieved via one of the three concurrency control models, namely, bulk synchronization processing (BSP), asynchronous processing, and synchronous processing. Among them, synchronous processing has the potential to achieve the best performance due to fine-grained parallelism, while ensuring the correctness and the convergence of the computation, if an effective concurrency control scheme is used. This paper explores the topological properties of the underlying graph to design and implement a highly effective concurrency control scheme for efficient synchronous processing in an in-memory graph analytical engine. Our design uses a novel hybrid approach that combines 2PL (two-phase locking) with OCC (optimistic concurrency control), for high degree and low degree vertices in a graph respectively. Our results show that the proposed hybrid synchronous scheduler has significantly outperformed other synchronous schedulers in existing graph analytical engines, as well as BSP and asynchronous schedulers.

Abstract:To hide the complexity of the underlying system, graph processing frameworks ask programmers to specify graph computations in user-defined functions (UDFs) of graph-oriented programming model. Due to the nature of distributed execution, current frameworks cannot precisely enforce the semantics of UDFs, leading to unnecessary computation and communication. It exemplifies a gap between programming model and runtime execution. This article proposes novel graph processing frameworks for distributed system and Processing-in-memory (PIM) architecture that precisely enforces loop-carried dependency; i.e., when a condition is satisfied by a neighbor, all following neighbors can be skipped. Our approach instruments the UDFs to express the loop-carried dependency, then the distributed execution framework enforces the precise semantics by performing dependency propagation dynamically. Enforcing loop-carried dependency requires the sequential processing of the neighbors of each vertex distributed in different nodes. We propose to circulant scheduling in the framework to allow different nodes to process disjoint sets of edges/vertices in parallel while satisfying the sequential requirement. The technique achieves an excellent trade-off between precise semantics and parallelism-the benefits of eliminating unnecessary computation and communication offset the reduced parallelism. We implement a new distributed graph processing framework SympleGraph, and two variants of runtime systems-GraphS and GraphSR-for PIM-based graph processing architecture, which significantly outperform the state-of-the-art.
Congra: Towards Efficient Processing of Concurrent Graph Queries on Shared-Memory Machines

Abstract:Parallel graph processing has been routinely used to solve problems in a wide range of real life applications today. Efficiently handling many concurrent graph processing queries in a multi-user environment is highly desirable as we enter a world full of edge device oriented services. Existing research, however, primarily focuses on processing a single, large graph dataset and leaves the efficient handling of multiple mid-sized graph queries an interesting yet challenging open problem. In this work, we investigate the management of multiple graph processing queries on shared-memory machines. We carefully analyze the performance of several graph algorithms and find some of them do not scale well with more CPU cores (more threads) while others have diminishing returns as the number of CPU cores grow. Further, we identify the trade-off relationship between the increasing cost of atomic operations and the growing available memory bandwidth with more CPU cores. Motivated by the above observations, we propose Congra, a dynamic graph scheduler that intelligently manages multiple concurrent graph queries for better system throughput and resource efficiency. Congra collects the memory bandwidth consumption and atomic operations characteristics of graph queries via offline profiling and decides which subset of CPU cores for the query to run, as long as the query is not blocked due to heavy resources contention. We implement Congra in C++ on top of the Ligra graph processing framework and test it with judiciously selected graph processing query combinations. Our results show the Congra improves query throughput by 60% compared to existing designs. It exhibits much better quality of service and readily supports a scale-out computing environment.
SympleGraph: Distributed Graph Processing with Precise Loop-Carried Dependency Guarantee.

The significant speedups in most graphs and algorithms indicate that the benefits of eliminating unnecessary computation and communication overshadow the reduced parallelism. Communication efficiency is further optimized by 1) selectively propagating dependency for large-degree vertices to increase net benefits; 2) double buffering to hide communication latency. In a 16-node cluster, SympleGraph outperforms the state-of-the-art system Gemini and D-Galois on average by 1.42× and 3.30×, and up to 2.30× and 7.76×, respectively. The communication reduction compared to Gemini is 40.95% on average and up to 67.48%.
GraphHP: A Hybrid Platform for Iterative Graph Processing.

Abstract:The Bulk Synchronous Parallel(BSP) computational model has emerged as the dominant distributed framework to build large-scale iterative graph processing systems. While its implementations(e.g., Pregel, Giraph, and Hama) achieve high scalability, frequent synchronization and communication among the workers can cause substantial parallel inefficiency. To help address this critical concern, this paper introduces the GraphHP(Graph Hybrid Processing) platform which inherits the friendly vertex-centric BSP programming interface and optimizes its synchronization and communication overhead. To achieve the goal, we first propose a hybrid execution model which differentiates between the computations within a graph partition and across the partitions, and decouples the computations within a partition from distributed synchronization and communication. By implementing the computations within a partition by pseudo-superstep iteration in memory, the hybrid execution model can effectively reduce synchronization and communication overhead while not requiring heavy scheduling overhead or graph-centric sequential algorithms. We then demonstrate how the hybrid execution model can be easily implemented within the BSP abstraction to preserve its simple programming interface. Finally, we evaluate our implementation of the GraphHP platform on classical BSP applications and show that it performs significantly better than the state-of-the-art BSP implementations. Our GraphHP implementation is based on Hama, but can easily generalize to other BSP platforms.

Abstract:Popular distributed graph processing frameworks, such as Pregel and GraphLab, are based on the vertex-centric computation model, where users write their customized Compute function for each vertex to process the data iteratively. Vertices are evenly partitioned among the compute nodes, and the granularity of parallelism of the graph algorithm is normally tuned by adjusting the number of compute nodes. Vertex-centric model splits the computation into phases. Inside one specific phase, the computation proceeds as an embarrassingly parallel process, because no communication between compute nodes incurs. By default, current graph engine only handles one iteration of the algorithm in a phase. However, in this paper, we find that we can also tune the granularity of parallelism, by aggregating the computation of multiple iterations into one phase, which has a significant impact on the performance of the graph algorithm. In the ideal case, if all computations are handled in one phase, the whole algorithm turns into an embarrassingly parallel algorithm and the benefit of parallelism is maximized. Based on this observation, we propose two approaches, a function-based approach and a parameter-based approach, to automatically transform a Pregel algorithm into a new one with tunable granularity of parallelism. We study the cost of such transformation and the trade-off between the granularity of parallelism and the performance. We provide a new direction to tune the performance of parallel algorithms. Finally, the approaches are implemented in our graph processing system, N2, and we illustrate their performance using popular graph algorithms.
Distributed PathGraph: A Cluster Centric Framework for Distributed Processing Graph

Abstract:Large scale graph processing represents an interesting challenge due to the characteristics of the graph structure. Generally, a distributed graph processing framework is a better choice for large graphs with billions of edges. However, traditional iterative computation models like BSP under-perform due to large communication overheads and slow iterative convergence in a distributed environment. Here, we present DistPathGraph, a distributed graph processing framework based on PathGraph. First, considering the difference between single machine and cluster, we describe a novel cluster based partitioning method that is different from PathGraph. Second, due to dependence of vertices and consistency of data replicas in different partitions, we present a scheme to control the order of vertices in the updating procedure. Finally, we design a message-packing strategy that improves communication congestion and the rate of iterative convergence. Generally, synchronous communication model controls the computation and communication steps by barrier, which induces more CPU idle time and communication congestion. Although asynchronous model can eliminate CPU idle in some sense, it may lead to inconsistency of vertices and require complex control logic. Comparing to two models, our strategy is a better compromise. We evaluate our graph processing framework against GraphLab. The experimental results validate that our partitioning method and communication strategy improve performance, and that our graph processing framework outperforms GraphLab by up to 6.53X.

Abstract:Distributed processing of large-scale graph data has many practical applications and has been widely studied. In recent years, a lot of distributed graph processing frameworks and algorithms have been proposed. While many efforts have been devoted to analyzing these, with most analyzing them based on programming models, less research focuses on understanding their challenges in distributed environments. Applying graph tasks to distributed environments is not easy, often facing numerous challenges through our analysis, including parallelism, load balancing, communication overhead, and bandwidth. In this paper, we provide an extensive overview of the current state-of-the-art in this field by outlining the challenges and solutions of distributed graph algorithms. We first conduct a systematic analysis of the inherent challenges in distributed graph processing, followed by presenting an overview of existing general solutions. Subsequently, we survey the challenges highlighted in recent distributed graph processing papers and the strategies adopted to address them. Finally, we discuss the current research trends and identify potential future opportunities.

Further, based on the survey, we have made classifications and comparisons. At last, we have presented the prospects of the possible development direction of concurrency bug debugging approaches.
GraphTune: an Efficient Dependency-Aware Substrate to Alleviate Irregularity in Concurrent Graph Processing

Abstract:With the increasing need for graph analysis, massive Concurrent iterative Graph Processing (CGP) jobs are usually performed on the common large-scale real-world graph. Although several solutions have been proposed, these CGP jobs are not coordinated with the consideration of the inherent dependencies in graph data driven by graph topology. As a result, they suffer from redundant and fragmented accesses of the same underlying graph dispersed over distributed platform, because the same graph is typically irregularly traversed by these jobs along different paths at the same time. In this work, we develop GraphTune , which can be integrated into existing distributed graph processing systems, such as D-Galois, Gemini, PowerGraph, and Chaos, to efficiently perform CGP jobs and enhance system throughput. The key component of GraphTune is a dependency-aware synchronous execution engine in conjunction with several optimization strategies based on the constructed cross-iteration dependency graph of chunks. Specifically, GraphTune transparently regularizes the processing behavior of the CGP jobs in a novel synchronous way and assigns the chunks of graph data to be handled by them based on the topological order of the dependency graph so as to maximize the performance. In this way, it can transform the irregular accesses of the chunks into more regular ones so that as many CGP jobs as possible can fully share the data accesses to the common graph. Meanwhile, it also efficiently synchronizes the communications launched by different CGP jobs based on the dependency graph to minimize the communication cost. We integrate it into four cutting-edge distributed graph processing systems and a popular out-of-core graph processing system to demonstrate the efficiency of GraphTune. Experimental results show that GraphTune improves the throughput of CGP jobs by 3.1∼6.2, 3.8∼8.5, 3.5∼10.8, 4.3∼12.4, and 3.8∼6.9 times over D-Galois, Gemini, PowerGraph, Chaos, and GraphChi, respectively.
Graph3S: A Simple, Speedy and Scalable Distributed Graph Processing System

Abstract: Graph is a ubiquitous structure in many domains. The rapidly increasing data volume calls for efficient and scalable graph data processing. In recent years, designing distributed graph processing systems has been an increasingly important area to fulfil the demands of processing big graphs in a distributed environment. Though a variety of distributed graph processing systems have been developed, very little attention has been paid to achieving a good combinational system performance in terms of usage simplicity, efficiency and scalability. To contribute to the study of distributed graph processing system, this work tries to fill this gap by designing a simple, speedy and scalable system. Our observation is that enforcing the communication flexibility of a system leads to the gains of both system efficiency and scalability as well as simple usage. We realize our idea in a system Graph3S and conduct extensive experiments with diverse algorithms over big graphs from different domains to test its performance. The results show that, besides simple usage, our system has outstanding performance over various graph algorithms and can even reach up to two orders of magnitude speedup over existing in-memory systems when applying to some algorithms. Also, its scalability is competitive to disk-based systems and even better when less machines are used.
Optimizing Declarative Parallel Distributed Graph Processing by Using Constraint Solvers.

Abstract:Vertex-centric graph processing is a promising approach for facilitating development of parallel distributed graph processing programs. Each vertex is regarded as a tiny thread and graph processing is described as cooperation among vertices. This approach resolves many issues in parallel distributed processing such as synchronization and load balancing. However, it is still difficult to develop efficient programs requiring careful problem-specific tuning. We present a method for automatically optimizing vertex-centric graph processing programs. The key is the use of constraint solvers to analyze the subtle properties of the programs. We focus on a functional vertex-centric graph processing language, Fregel, and show that quantifier elimination and SMT (Satisfiability Modulo Theories) are useful for optimizing Fregel programs. A preliminary experiment indicated that a modern SMT solver can perform optimization within a realistic time frame and that our method can significantly improve the performance of naively written declarative vertex-centric graph processing programs.
SPDebugger: A Fine-Grained Deterministic Debugger for Concurrency Code

Abstract:When debugging bugs, programmers often prepare test cases to reproduce buggy behaviours. However, for concurrent programs, test cases alone are typically insufficient to reproduce buggy behaviours, due to the nondeterminism of multi-threaded executions. In literature, various approaches have been proposed to reproduce buggy behaviours for concurrency bugs deterministically, but to the best of our knowledge, they are still limited. In particular, we have recognized three debugging scenarios from programming practice, but existing approaches can handle only one of the scenarios. In this paper, we propose a novel approach, called SPDebugger, that provides finer-grained thread controlling over test cases, programs under test, and even third party library code, to reproduce the pre-designed thread execution schedule. The evaluation shows that SPDebugger handles more debugging scenarios than the state-of-the-art tool, called IMUnit, with similar human effort.
CGraph: A Correlations-aware Approach for Efficient Concurrent Iterative Graph Processing

Abstract:With the fast growing of iterative graph analysis applications, the graph processing platform has to efficiently handle massive Concurrent iterative Graph Processing (CGP) jobs. Although it has been extensively studied to optimize the execution of a single job, existing solutions face high ratio of data access cost to computation for the CGP jobs due to significant cache interference and memory wall, which incurs low throughput. In this work, we observed that there are strong spatial and temporal correlations among the data accesses issued by different CGP jobs because these concurrently running jobs usually need to repeatedly traverse the shared graph structure for the iterative processing of each vertex. Based on this observation, this paper proposes a correlations-aware execution model, together with a core-subgraph based scheduling algorithm, to enable these CGP jobs to efficiently share the graph structure data in cache/memory and their accesses by fully exploiting such correlations. It is able to achieve the efficient execution of the CGP jobs by effectively reducing their average ratio of data access cost to computation and therefore delivers a much higher throughput. In order to demonstrate the efficiency of the proposed approaches, a system called CGraph is developed and extensive experiments have been conducted. The experimental results show that CGraph improves the throughput of the CGP jobs by up to 2.31 times in comparison with the existing solutions.

Abstract:With the globalization of manufacturing and product development activities, the need for collaborative environment supporting a wide range of engineering design and product performance evaluation becomes much more important. One of the most critical problems involved in the integration of CAE capabilities in the distributed and collaborative product development environment is concurrency management. The problem is challenging as concurrency in collaboration process, dependable computing tasks and engineering data is often highly complex. In this study, a distributed and collaborative CAD/CAE framework, which is to provide reliable support to CAD and CAE sessions participated by designers from geographically dispersed locations, is presented. The concurrency problem in collaborative CAD/CAE environment is discussed. A multi-thread synchronizing scheme for collaboration synchronization is proposed to realize efficient real-time interaction for both CAD and CAE processes.
Superscalar Communication: A Runtime Optimization for Distributed Applications

Abstract:Building distributed applications is difficult mostly because of concurrency management. Existing approaches primarily include events and threads. Researchers and developers have been debating for decades to prove which is superior. Although the conclusion is far from obvious, this long debate clearly shows that neither of them is perfect. One of the problems is that they are both complex and error-prone. Both events and threads need the programmers to explicitly manage concurrencies, and we believe it is just the source of difficulties. In this paper, we propose a novel approach—superscalar communication, in which concurrencies are automatically managed by the runtime system. It dynamically analyzes the programs to discover potential concurrency opportunities; and it dynamically schedules the communication and the computation tasks, resulting in automatic concurrent execution. This approach is inspired by the idea of superscalar technology in modern microprocessors, which dynamically exploits instruction-level parallelism. However, hardware superscalar algorithms do not fit software in many aspects, thus we have to design a new scheme completely from scratch. Superscalar communication is a runtime extension with no modification to the language, compiler or byte code, so it is good at backward compatibility. Superscalar communication is likely to begin a brand new research area in systems software, which is characterized by dynamic optimization for networking programs.
