Abstract:Massive Open Online Courses (MOOCs) are playing a key role in improving educational ways. Abundant learning resources make it difficult for online users to find suitable learning content. The current personalized service in the field of online education relies more on course recommendations. However, coarse-grained recommendations cannot help users discover the defects of their knowledge network effectively. In this paper, we propose a Knowledge-Aware Meta-Concept (KAMC) framework to provide fine-grained recommendation services. We innovatively incorporate Knowledge Graph (KG) into the field of educational recommendation to provide abundant auxiliary information. However, simply combining knowledge graphs with educational recommender systems cannot improve the performance of existing recommendation models, and may even weaken the performance of the models. Because the modeled KG ignores the enhancements on the user side and only considers the enhancements on the item side. We further propose to enrich the semantic representation of users with collaborative information in user-item interactions, and at the same time enrich the semantic representation of items with information in KG. Furthermore, to provide users with more accurate and fine-grained personalized recommendation services, we propose a user-based attention mechanism to capture users’ fine-grained semantic information. Our method is experimentally validated on three real-world datasets. In the three datasets, KAMC’s AUC evaluation index is 6.2% , 6.9% , and 2.2% higher than the latest baseline method (KGAN), respectively. Experimental results show that the KAMC method outperforms the current state-of-the-art baseline methods.
MOOCon: A Framework for Semi-supervised Concept Extraction from MOOC Content

Abstract:Recent years have witnessed the rapid development of Massive Open Online Courses (MOOCs). MOOC platforms not only offer a one-stop learning setting, but also aggregate a large number of courses with various kinds of textual content, e.g. video subtitles, quizzes and forum content. MOOCs are also regarded as a large-scale ‘knowledge base’ which covers various domains. However, all the contents generated by instructors and learners are unstructured. In order to process the data to be structured for further knowledge management and mining, the first step could be concept extraction. In this paper, we expect to utilize human knowledge through labeling data, and propose a framework for concept extraction based on machine learning methods. The framework is flexible to support semi-supervised learning, in order to alleviate human effort of labeling training data. Also course-agnostic features are designed for modeling cross-domain data. Experimental results demonstrate that only 10% labeled data can lead to acceptable performance, and the semi-supervised learning method is comparable to the supervised version under the consistent framework. We find the textual contents of various forms, i.e. subtitles, PPTs and questions, should be separately processed due to their formal difference. At last we evaluate a new task: identifying needs of concept comprehension. Our framework can work well in doing identification on forum content while learning a model from subtitles.

Abstract:Massive Open Online Courses (MOOCs), offering a new way to study online, are revolutionizing education. One challenging issue in MOOCs is how to design effective and fine-grained course concepts such that students with different backgrounds can grasp the essence of the course. In this paper, we conduct a systematic investigation of the problem of course concept extraction for MOOCs. We propose to learn latent representations for candidate concepts via an embedding-based method. Moreover, we develop a graph-based propagation algorithm to rank the candidate concepts based on the learned representations. We evaluate the proposed method using different courses from XuetangX and Coursera. Experimental results show that our method significantly outperforms all the alternative methods (+0.013-0.318 in terms of R-precision; p<<0.01, t-test).

Abstract:Massive Open Online Courses(MOOCs) provide convenient access to knowledge for learners all over the world. Concept Extraction is a basic requirement in MOOCs. However, textual content in MOOCs, such as video subtitles and quizzes, are generally presented as semi-structured or unstructured format. Thus it is hard to extract important concepts with simple methods from MOOCs. In this paper, we design a graph-based propagation method to solve the concept extraction problem. Our method utilize textual and structured data on Wikipedia, to generate implicit and explicit representation for concepts respectively. Experiments show that our method outperforms alternative methods on Chinese dataset(+0.054-0.062 in terms of MAP).

Abstract:As Massive Open Online Courses (MOOCs) become increasingly popular, it is promising to automatically provide extracurricular knowledge for MOOC users. Suffering from semantic drifts and lack of knowledge guidance, existing methods can not effectively expand course concepts in complex MOOC environments. In this paper, we first build a novel boundary during searching for new concepts via external knowledge base and then utilize heterogeneous features to verify the high-quality results. In addition, to involve human efforts in our model, we design an interactive optimization mechanism based on a game. Our experiments on the four datasets from Coursera and XuetangX show that the proposed method achieves significant improvements(+0.19 by MAP) over existing methods. Abstract:With the rapid growth of Massive Open Online Courses (MOOCs), it is expensive and time-consuming to extract high-quality knowledgeable concepts taught in the course by human effort to help learners grasp the essence of the course.In this paper, we propose to automatically extract course concepts using distant supervision to eliminate the heavy work of human annotations, which generates labels by matching them with an easily accessed dictionary.However, this matching process suffers from severe noisy and incomplete annotations because of the limited dictionary and diverse MOOCs.To tackle these challenges, we present a novel three-stage framework DS-MOCE, which leverages the power of pretrained language models explicitly and implicitly and employs discipline-embedding models with a self-train strategy based on label generation refinement across different domains.We also provide an expert-labeled dataset spanning 20 academic disciplines.Experimental results demonstrate the superiority of DS-MOCE over the state-of-the-art distantly supervised methods (with 7% absolute F1 score improvement).Code and data are now available at https: //github.com/THU-KEG/MOOC-NER.

Abstract:The emerging Semantic Web has facilitated the incorporation of various large-scale on-line ontologies and semantic-based applications; howbeit Web ontologies are due to their complex nature far from being a commodity and make user exploration run into a number of difficulties. Concept maps that provide visual languages for organizing and representing knowledge may complement Web ontologies in several aspects to support efficient knowledge reuse. In this paper, we propose, on top of the Semantic Web technology, an interactive visual model that extends Web ontology with concept map for exploring Web ontologies. We propose several algorithms from the point of view of the graph theory to analyze and uncover some underlying characteristics, to enhance Web ontology exploration in some novel aspects.

Abstract:With the prevalence of web-based learning, the application of concept mapping, as a powerful diagnostic and instructional tool, has been widely exploited in both education and computer science. In recent years, several methods have been presented to automatically construct concept map that achieved encouraging results, while ignoring some critical issues when applied in actual E-learning system. In this paper, we propose a practical approach for constructing concept map, which is adapted to the dynamic character of a real system. Moreover, we apply fuzzy set theory and fuzzy reasoning basis on fuzzy rules for similarity degree between two concepts, to find direct prerequisite relationship among concepts. It provides a useful way to improve accuracy and reduce complexity of the concept map.

Abstract:In this article, we study knowledge concept recommendation in Massive Open Online Courses (MOOCs) in an explainable manner. Knowledge concepts, composing course units (e.g., videos) in MOOCs, refer to topics and skills that students are expected to master. Compared to traditional course recommendation in MOOCs, knowledge concepts recommendation has drawn more attention because students’ interests over knowledge concepts can better revealstudents’ real intention in a more refined granularity. However, there are three unique challenges in knowledge concept recommendation: (1) How to design an appropriate data structure to capture complex relationships between knowledge concepts, course units, and other participants (e.g., students, teachers)? (2) How to model interactions between students and knowledge concepts? (3) How to make explainable recommendation results to students? To tackle these challenges, we formulate the knowledge concept recommendation as a reinforcement learning task integrated with MOOC knowledge graph (KG). Specifically, we first construct MOOC KG as the environment to capture all the relationships and behavioral histories by considering all the entities (e.g., students, teachers, videos, courses, and knowledge concepts) on the MOOC provider. Then, to model the interactions between students and knowledge concepts, we train an agent to mimic students’ learning behavioral patterns facing the complex environment. Moreover, to provide explainable recommendation results, we generate recommended knowledge concepts in the format of a path from MOOC KG to indicate semantic reasons. Finally, we conduct extensive experiments on a real-world MOOC dataset to demonstrate the effectiveness of our proposed method.

Abstract:Massive Open Online Courses (MOOCs) have gained tremendous popularity in the last few years. Discussion forums are a common element in MOOCs. Previously, Numerous studies have been undertaken on the potential role that discussion forums play in education. However, the existing works don’t effectively mine and analyze the rich text information of the forums associated with learner performances. In this work, we propose a hybrid method to mine learner roles based on MOOC discussion forums and to jointly evaluate the quality of learning with other learning activities. We pay more attention to extracting semantic features of posts and comments in forums, which help to promote the performance prediction. We evaluate the performance of our method based on the Coursera platform. Experiments show that our approach can improve the performance compared to existing works on these tasks.
A Top-down Graph-based Tool for Modeling Classical Semantic Maps: A Crosslinguistic Case Study of Supplementary Adverbs

Abstract:Semantic map models (SMMs) construct a network-like conceptual space from cross-linguistic instances or forms, based on the connectivity hypothesis. This approach has been widely used to represent similarity and entailment relationships in cross-linguistic concept comparisons. However, most SMMs are manually built by human experts using bottom-up procedures, which are often labor-intensive and time-consuming. In this paper, we propose a novel graph-based algorithm that automatically generates conceptual spaces and SMMs in a top-down manner. The algorithm begins by creating a dense graph, which is subsequently pruned into maximum spanning trees, selected according to metrics we propose. These evaluation metrics include both intrinsic and extrinsic measures, considering factors such as network structure and the trade-off between precision and coverage. A case study on cross-linguistic supplementary adverbs demonstrates the effectiveness and efficiency of our model compared to human annotations and other automated methods. Abstract:The prosperity of massive open online courses provides fodder for plentiful research efforts on adaptive learning. However, current open-access educational datasets are still far from sufficient to meet the need for various topics of adaptive learning. Existing released datasets often cover only small-scale data, lack fine-grained knowledge concepts. They are even difficult to curate and supplement due to platform limitations. In this work, we construct MOOCCubeX, a large, knowledge-centered repository consisting of 4, 216 courses, 230, 263 videos, 358, 265 exercises, 637, 572 fine-grained concepts and over 296 million behavioral data of 3, 330, 294 students, for supporting the research topics on adaptive learning in MOOCs. Licensed by XuetangX, one of the largest MOOC websites in China, we obtain abundant and diverse course resources and student behavioral data and are permitted to make subsequent periodic updates. We propose a framework to accomplish data processing, weakly supervised fine-grained concept graph mining, and data curation to improve usability and richness. Based on the fine-grained concepts, we re-organize the data from the knowledge perspective and acquire more external learning resources from the web. Abstract:Purpose Recent years have witnessed the rapid development of massive open online courses (MOOCs). With more and more courses being produced by instructors and being participated by learners all over the world, unprecedented massive educational resources are aggregated. The educational resources include videos, subtitles, lecture notes, quizzes, etc., on the teaching side, and forum contents, Wiki, log of learning behavior, log of homework, etc., on the learning side. However, the data are both unstructured and diverse. To facilitate knowledge management and mining on MOOCs, extracting keywords from the resources is important. This paper aims to adapt the state-of-the-art techniques to MOOC settings and evaluate the effectiveness on real data. In terms of practice, this paper also tries to answer the questions for the first time that to what extend can the MOOC resources support keyword extraction models, and how many human efforts are required to make the models work well. Design/methodology/approach Based on which side generates the data, i.e instructors or learners, the data are classified to teaching resources and learning resources, respectively. The approach used on teaching resources is based on machine learning models with labels, while the approach used on learning resources is based on graph model without labels. Findings From the teaching resources, the methods used by the authors can accurately extract keywords with only 10 per cent labeled data. The authors find a characteristic of the data that the resources of various forms, e.g. subtitles and PPTs, should be separately considered because they have the different model ability. From the learning resources, the keywords extracted from MOOC forums are not as domain-specific as those extracted from teaching resources, but they can reflect the topics which are lively discussed in forums. Then instructors can get feedback from the indication. The authors implement two applications with the extracted keywords: generating concept map and generating learning path. The visual demos show they have the potential to improve learning efficiency when they are integrated into a real MOOC platform. Research limitations/implications Conducting keyword extraction on MOOC resources is quite difficult because teaching resources are hard to be obtained due to copyrights. Also, getting labeled data is tough because usually expertise of the corresponding domain is required. Practical implications The experiment results support that MOOC resources are good enough for building models of keyword extraction, and an acceptable balance between human efforts and model accuracy can be achieved. Originality/value This paper presents a pioneer study on keyword extraction on MOOC resources and obtains some new findings.

Abstract:Since its introduction in 2011, there have been over 4000 MOOCs on various subjects on the Web, serving over 35 million learners. MOOCs have shown the ability to democratize knowledge dissemination and bring the best education in the world to every learner. However, the disparate distances between participants, the size of the learner population, and the heterogeneity of the learners' backgrounds make it extremely difficult for instructors to interact with the learners in a timely manner, which adversely affects learning experience. To address the challenges, in this thesis, we propose a framework: educational content linking. By linking and organizing pieces of learning content scattered in various course materials into an easily accessible structure, we hypothesize that this framework can provide learners guidance and improve content navigation. Since most instruction and knowledge acquisition in MOOCs takes place when learners are surveying course materials, better content navigation may help learners find supporting information to resolve their confusion and thus improve learning outcome and experience. To support our conjecture, we present end-to-end studies to investigate our framework around two research questions: 1) can manually generated linking improve learning? 2) can learning content be generated with machine learning methods? For studying the first question, we built an interface that present learning materials and visualize the linking among them simultaneously. We found the interface enables users to search for desired course materials more efficiently, and retain more concepts more readily. For the second question, we propose an automatic content linking algorithm based on conditional random fields. We demonstrate that automatically generated linking can still lead to better learning, although the magnitude of the improvement over the unlinked interface is smaller.
Research on a New Automatic Generation Algorithm of Concept Map Based on Text Clustering and Association Rules Mining

Abstract:AbstractAs an important teaching tool of visualization, the concept map has become a hot spot in the field of smart education. The traditional concept map generation algorithm is hard to guarantee the construction process and quality because of the huge amount of work and the great influence of the expert experience. A TC-ARM algorithm for automatic generation of hybrid concept map based on text clustering and association rules mining is proposed. This algorithm takes full account of the attributes of the relationship between concepts, uses text clustering technology to replace the relationship between artificial mining concepts and test questions, combines association rules mining methods to generate the concept maps, and introduces consistency of answer record parameter to improve the efficiency of concept map generation. The experimental results show that the TC-ARM algorithm can automatically and rapidly construct the concept map, which not only reduces the impact of outside experts, but also dynamically adjusts the concept map based on the basic data. The concept map generated by the TC-ARM algorithm expresses the relationship between the concepts and the degree of closeness through the relationship pairs and relationship strength, and can clearly show the structural relationship between concepts, provide instructional optimization guidance for knowledge visualization.

Abstract:Recent advances in Web and information technologies have resulted in many e-learning resources. There is an emerging requirement to manage and reuse relevant resources together to achieve on-demand e-learning in the Web. Ontologies have become a key technology for enabling semantic-driven resource management. We argue that to meet the requirements of semantic-based resource management for Web-based e-learning, one should go beyond using domain ontologies statically. In this paper, we provide a semantic mapping mechanism to integrate e-learning databases by using ontology semantics. Heterogeneous e-learning databases can be integrated under a mediated ontology. Taking into account the locality of resource reuse, we propose to represent context-specific portions from the whole ontology as subontologies. We present a subontology-based approach for resource reuse by using an evolutionary algorithm. We also conduct simulation experiments to evaluate the approach with a traditional Chinese medicine e-learning scenario and obtain promising results.

Abstract:For an innovation producing education, MOOC (Massive Open Online Course) platforms offer a plethora of learning resources and pedagogical activities to support the university’s 4.0 new era and the lifelong learning movement. Nevertheless, the rapid advances in learning technologies imply the need for personalized guidance for learners and adapted learning materials. In this paper we seek to enhance the MOOC learner experience by providing a semantic recommender system for the diversity and abundance of MOOCs available for learners. Firstly, the paper analyses the state of the art of the semantic recommendation approach in a distance learning context. Then it describes the proposed MOOC recommendation system that uses the ontological representation of the learner model and MOOCs content to make its intelligent suggestions. Finally, we explore the development phases of the semantic MOOC recommendation system to define the implications for the progress of our research.

Abstract:Many machine learning models have been built to tackle information overload issues on Massive Open Online Courses (MOOC) platforms. These models rely on learning powerful representations of MOOC entities. However, they suffer from the problem of scarce expert label data. To overcome this problem, we propose to learn pre-trained representations of MOOC entities using abundant unlabeled data from the structure of MOOCs which can directly be applied to the downstream tasks. While existing pre-training methods have been successful in NLP areas as they learn powerful textual representation, their models do not leverage the richer information about MOOC entities. This richer information includes the graph relationship between the lectures, concepts, and courses along with the domain knowledge about the complexity of a concept. We develop MOOCRep, a novel method based on Transformer language model trained with two pre-training objectives : 1) graph-based objective to capture the powerful signal of entities and relations that exist in the graph, and 2) domain-oriented objective to effectively incorporate the complexity level of concepts. Our experiments reveal that MOOCRep's embeddings outperform state-of-the-art representation learning methods on two tasks important for education community, concept pre-requisite prediction and lecture recommendation.
