Abstract:Data-driven methods [1] are transforming the engineering, physical, and biological sciences. Indeed, innovative uses of machine learning [2–4], dimensionality reduction [1–4], equation-free methods [5–7], sparse sensing [8–11], and/or network characterization techniques are allowing for significant advances in engineering designs for the prediction and control of highly complex, often networked, systems. Integrating together one or more of the aforementioned methodologies often provides transformative analytical tools and algorithms for characterizing the underlying, typically low-dimensional, dynamics of the complex system. Despite their myriad successes, many of these innovative mathematical strategies have yet to be applied to a wide range of engineering systems. Of particular interest in this manuscript is the use of modern data methods for building self-tuning optical systems such as mode-locked lasers [12–16]. Thus, we demonstrate how machine learning strategies coupled with sparse sensing can provide a transformative paradigm for enacting adaptive and robust control laws for self-tuning complex systems. To demonstrate how data-driven modeling strategies can be applied generally in complex systems, a case study of mode-locked fiber lasers is conducted. Although more than two decades in development, such fiber lasers have yet to realize an adaptive, robust, and self-tuning control schemes capable of revolutionizing both commercial and academic sectors of ultrafast science. Abstract:Mode-locked fiber lasers based on nonlinear polarization rotation (NPR) have been widely applied due to the simple setup, high performance and rich nonlinear dynamics. However, temperature, vibration, and stress can easily disrupt the optimized mode-locked state. To address this problem, automatic mode-locked lasers using different self-tuning algorithms are proposed in recent years. However, it is relatively difficult to verify and optimize the performance of self-tuning algorithm since the use of actual laser platforms, which hinders the development of intelligent mode-locked fiber laser. In this paper, we demonstrate a simulation platform for NPR mode-locked fiber lasers by using coupled Ginzburg-Landau equation and Jones matrix, which makes the optimization of intelligent self-tuning algorithm easier. As a proof-of-principle demonstration, genetic algorithm and human-like algorithm are implemented to prove the ability of comparing different self-tuning algorithms.
Self-optimizing additive pulse mode-locked fiber laser: wavelength tuning and selective operation in continuous-wave or mode-locked regime

Abstract:Additive pulsed-mode mode-locked fiber lasers are known for their wide range of operating states, which can be achieved by tuning the artificial saturable absorber with built-in polarization controllers. We have equipped our laser with three motorized polarization controllers and online monitoring. We recorded three dimensional high-resolution maps of the oscillation states by stepping trough all possible polarization controller settings. In addition, we demonstrate the single and multi-objective optimization by a genetic algorithm of the fiber laser towards a desired operating state. To the best of our knowledge this is the first demonstration of multi-objective optimization of a fiber laser. Doing so, we can selectively operate the cavity in pulsed and continuous-wave mode and tune the wavelength of the laser emission by more than 55 nm. The high wavelength tunability is possible because the polarization controllers and the inline-polarizer act as a tunable birefringent filter.

Abstract:Increasing complexity of modern laser systems, mostly originated from the nonlinear dynamics of radiation, makes control of their operation more and more challenging, calling for development of new approaches in laser engineering. Machine learning methods, providing proven tools for identification, control, and data analytics of various complex systems, have been recently applied to mode-locked fiber lasers with the special focus on three key areas: self-starting, system optimization and characterization. However, the development of the machine learning algorithms for a particular laser system, while being an interesting research problem, is a demanding task requiring arduous efforts and tuning a large number of hyper-parameters in the laboratory arrangements. It is not obvious that this learning can be smoothly transferred to systems that differ from the specific laser used for the algorithm development by design or by varying environmental parameters. Here we demonstrate that a deep reinforcement learning (DRL) approach, based on trials and errors and sequential decisions, can be successfully used for control of the generation of dissipative solitons in mode-locked fiber laser system. We have shown the capability of deep Q-learning algorithm to generalize knowledge about the laser system in order to find conditions for stable pulse generation. Region of stable generation was transformed by changing the pumping power of the laser cavity, while tunable spectral filter was used as a control tool. Deep Q-learning algorithm is suited to learn the trajectory of adjusting spectral filter parameters to stable pulsed regime relying on the state of output radiation. Our results confirm the potential of deep reinforcement learning algorithm to control a nonlinear laser system with a feed-back. We also demonstrate that fiber mode-locked laser systems generating data at high speed present a fruitful photonic test-beds for various machine learning concepts based on large datasets.

Abstract:Recent years have witnessed growing research interest in dual-wavelength mode-locked fiber lasers for their pivotal role in diverse applications and the exploration of nonlinear dynamics. Despite notable progress in their development, achieving reliable mode-locked dual-wavelength operation typically necessitates intricate manual adjustments of the cavity's polarization components. In this article, we present the realization of automatic mode-locking in a dual-wavelength soliton fiber laser. To provide guidance for the algorithm design, we systematically investigated the impact of polarization configurations and initial states on the laser's operation through numerical simulations and linear scan experiments. The results indicate that operational regimes can be finely adjusted around the wave plate position supporting the mode-locked dual-wavelength solution. Furthermore, the laser exhibits multiple stable states at the mode-locked dual-wavelength point, with critical dependence on the initial conditions. Accordingly, we developed a two-stage genetic algorithm that was demonstrated to be effective for realizing automatic dual-wavelength mode-locking. To further improve the performance of the algorithm, a feedforward neural network was trained and integrated into the algorithm, enabling accurate identification of the dual-wavelength states. This study provides valuable insights into understanding how polarization configurations and initial conditions impact the operational regimes of dual-wavelength mode-locked fiber lasers. The algorithm developed can be extended to optimize other systems with multiple stable states supported at the same parameter point.

Classification of birefringence in mode-locked fiber lasers using machine learning and sparse representation.

Abstract:It has been observed that changes in the birefringence, which are difficult or impossible to directly measure, can significantly affect mode-locking in a fiber laser. In this work we develop techniques to estimate the effective birefringence by comparing a test measurement of a given objective function against a learned library. In particular, a toroidal search algorithm is applied to the laser cavity for various birefringence values by varying the waveplate and polarizer angles at incommensurate angular frequencies, thus producing a time-series of the objective function. The resulting time series, which is converted to a spectrogram and then dimensionally reduced with a singular value decomposition, is then labelled with the corresponding effective birefringence and concatenated into a library of modes. A sparse search algorithm (L-1-norm optimization) is then applied to a test measurement in order to classify the birefringence of the fiber laser. Simulations show that the sparse search algorithm performs very well in recognizing cavity birefringence even in the presence of noise and/or noisy measurements. Once classified, the wave plates and polarizers can be adjusted using servo-control motors to the optimal positions obtained from the toroidal search. The result is an efficient, self-tuning laser. Abstract:Fiber mode-locked lasers are nonlinear optical systems that provide ultrashort pulses at high repetition rates. However, adjusting the cavity parameters is often a challenging task due to the intrinsic multistability of a laser system. Depending on the adjustment of the cavity parameters, the optical output may vary significantly, including Q-switching, single and multipulse, and harmonic mode-locked regimes. In this study, we demonstrate an experimental implementation of the Soft Actor–Critic algorithm for generating a harmonic mode-locked regime inside a state-of-the-art fiber laser with an ion-gated nanotube saturable absorber. The algorithm employs nontrivial strategies to achieve a guaranteed harmonic mode-locked regime with the highest order by effectively managing the pumping power of a laser system and the nonlinear transmission of a nanotube absorber. Our results demonstrate a robust and feasible machine-learning–based approach toward an automatic system for adjusting nonlinear optical systems with the presence of multistability phenomena.

Investigation of Dissipative Solitons in an Er-doped Fiber Laser Through Machine-Learning Online Optimization Based on the Gaussian Process

Abstract:We have applied a machine-learning online optimization method based on the Gaussian process to the numerical modeling of dissipative solitons in an Er-doped and nonlinear polarization rotation mode-locked fiber laser. Three types of dissipative solitons are achieved both experimentally and numerically in the negative, near-zero, and positive net cavity dispersion regions. Corresponding optimum cavity parameters in simulation can be determined quickly and precisely via optimization. The optimization goal is the high similarity between the experimental results and the simulation results, which is calculated by the sum of Fréchet distance of the normalized spectral waveforms and autocorrelation traces. In numerical analyses, the characteristics of the output pulse in different dispersion conditions, the pulse dynamics inside the laser cavity, and the initial process of mode-locking are also investigated. Our results demonstrate the effectiveness and universality of machine-learning online optimization based on the Gaussian process method in the optimization process of fiber laser modeling, which can further provide more insights and extend large-scale potential applications of machine-learning algorithms in fiber lasers.
Machine Learning Method for Calculating Mode-Locking Performance of Linear Cavity Fiber Lasers

Abstract:As a commonly used pulse light source, fiber mode-locked lasers are widely used in communication, frequency comb, nonlinear optics and other fields. Although people can accurately predict and analyze the performance of mode-locked pulse with given parameters of fiber laser by existing theories and calculation methods, it is difficult to analyze the mode-locked performance of fiber laser with multi-parameter changes by traditional methods. In this paper, we use machine learning technology to put forward a new view on this problem. Firstly, we use an artificial neural network (ANN) to judge whether a small noise pulse can evolve into a stable mode-locked state in the linear cavity fiber laser. Then, the time domain function of sample pulse is expanded by Fourier series. We use the Fourier coefficients as the network output and train another ANN that can predict the pulse shape quickly and accurately. Finally, we demonstrate how to use the genetic algorithm and the trained network to compute the parameters of the fiber laser when the given pulse width is known. The authors believe that the theoretical ideas and computational models presented in this work have great potential in the dynamics research and fabrication of fiber lasers.

Abstract:With the development of software-defined networking and coherent transmission, to name only a couple of emerging technical and technological areas, optical networks have rapidly expanded during the past few years. To handle with the enormous increment, several sections of optical transmission networks have been addressed via machine learning. Techniques such as support vector machine and KNN algorithms are widely used in fiber-induced nonlinear mitigation, which can cause enormous financial loses if the problem is not solved properly. Optical performance monitoring is another essential area in optical networks, which often adopts multitasking, while failure management, where anomaly detection takes place, rely on both supervised and unsupervised learning methods. The overview includes a brief synopsis of four types of learning methods, including supervised learning, unsupervised learning, semi-supervised learning and reinforcement, as well as the most recent advancements in methodologies used in optical fibre communication. At the end of the analysis, it is demonstrated that ML algorithms are selected based on the challenges present and we have to consider multiple factors when choosing a suitable algorithm. The combination of the two fields brings prosperity to each other.

Abstract:The diverse applications of mode-locked fiber lasers (MLFLs) raise various demands on the output of the laser, including the pulse duration, energy, and shape. Simulation is an excellent method to guide the design and construction of an MLFL for on-demand laser output. Traditional simulation of an MLFL uses the split-step Fourier method (SSFM) to solve the nonlinear Schrödinger (NLS) equation, which suffers from high computational complexity. As a result, the inverse design of MLFLs via the traditional SSFM-based simulation method relies on the design experience. Here, a completely data-driven approach for the inverse design of MLFLs is proposed, which significantly reduces the computational complexity and achieves a fast automatic inverse design of MLFLs. We utilize a recurrent neural network to realize fast and accurate MLFL modeling, then the desired cavity settings meeting the output demands are searched via a deep-reinforcement learning algorithm. The results prove that the data-driven method enables the accurate inverse design of an MLFL to produce a preset target femtosecond pulse with a certain duration and pulse energy. In addition, the cavity settings generating soliton molecules with different target separations can also be located via the data-driven inverse design. With the GPU acceleration, the time consumption of the data-driven inverse design of an MLFL is less than 1.3 hours. The proposed data-driven approach is applicable to guide the inverse design of an MLFL to meet the different demands of various applications.
Intelligent programmable mode-locked fiber laser with a human-like algorithm

Abstract:Nonlinear polarization evolution-based passively mode-locked fiber lasers with ultrafast and high peak power pulses are a powerful tool for engineering applications and scientific research. However, their sensitivity to polarization limits their widespread application. To address this, automatic mode-locking immune to environmental disturbances is gaining attention. Here, we experimentally demonstrate the first intelligent programmable mode-locked fiber laser enabled by our proposed human-like algorithm, combining the human approach with machine speed, computing capability, and precision. The laser is capable of automatically locking onto multiple operation regimes, such as fundamental mode-locking, harmonic mode-locking, Q -switching, and even Q -switched mode-locking without physically altering its structure. The shortest initial mode-locking time and recovery time from detachment are only 0.22 s and 14.8 ms, respectively, which are the record values to date. We believe this intelligent laser with superior performance can find practical applications in engineering and provide infinite possibilities for scientific research. © 2019 Optical Society of America under the terms of the OSA Open Access Publishing Agreement

Abstract:To improve the environmental stability and self-starting ability, researchers have developed the nonlinear optical-loop mirror and nonlinear amplifying-loop mirror (NALM) mode-locking technologies. The developing process of these technologies can be summarized as the following three phases: non-polarization-maintaining (PM) structures with polarization controllers, PM figure-of-8 cavity structures with dual-gain, and PM figure-of-9 cavity structures with a phase shifter. Among these, the newly invented figure-of-9 NALM mode-locked fiber laser is particularly advantageous owing to its easy self-starting ability, long-term stability, concise structure, and cost-effectiveness. Such a mode-locked fiber laser is increasingly employed in applications such as optical frequency combs, generation of THz radiation, and advanced material micromachining.

Abstract:We theoretically demonstrate that in a laser cavity mode-locked by nonlinear polarization rotation (NPR) using sets of waveplates and passive polarizer, the energy performance can be significantly increased by incorporating multiple NPR filters. The NPR filters are engineered so as to mitigate the multi-pulsing instability in the laser cavity which is responsible for limiting the single pulse per round trip energy in a myriad of mode-locked cavities. Engineering of the NPR filters for performance is accomplished by implementing a genetic algorithm that is capable of systematically identifying viable and optimal NPR settings in a vast parameter space. Our study shows that five NPR filters can increase the cavity energy by approximately a factor of five, with additional NPRs contributing little or no enhancements beyond this. With the advent and demonstration of electronic controls for waveplates and polarizers, the analysis suggests a general design and engineering principle that can potentially close the order of magnitude energy gap between fiber based mode-locked lasers and their solid state counterparts. Machine-learning Iterative Optimization for All Polarization-Maintaining Linear Cavity Er:fiber Laser.

Abstract:All polarization-maintaining (PM) linear cavity mode-locked fiber lasers are promising ultrafast laser sources due to their compactness and environmental robustness. Here, we demonstrate a linear cavity fiber laser with all-PM configuration experimentally and investigate the mode-locking formation of the laser using a machine-learning iterative optimization method based on the Gaussian process. The optimization algorithm can converge rapidly after only 30 runs. Using the optimized parameters, we simulate the generation of mode-locked pulses from noise. The output spectrum and pulse energy are highly consistent with the experiment. Furthermore, we describe the intracavity dynamic evolution under group velocity mismatch. We then show that the pulse trapping induced by cross-phase modulation leads to the overcompensated time synchronization between the orthogonally polarized components.
Controlling spatiotemporal nonlinearities in multimode fibers with deep neural networks

Abstract:Spatiotemporal nonlinear interactions in multimode fibers are of interest for beam shaping and frequency conversion by exploiting the nonlinear propagation of different pump regimes from quasi-continuous wave to ultrashort pulses centered around visible to infrared pump wavelengths. The nonlinear effects in multi-mode fibers depend strongly on the excitation condition, however relatively little work has been reported on this subject. Here, we present the first machine learning approach to learn and control the nonlinear frequency conversion inside multimode fibers by tailoring the excitation condition via deep neural networks. Trained with experimental data, deep neural networks are adapted to learn the relation between the spatial beam profile of the pump pulse and the spectrum generation. For different user-defined target spectra, network-suggested beam shapes are applied and control over the cascaded Raman scattering and supercontinuum generation processes are achieved. Our results present a novel method to tune the spectra of a broadband source.

Self-Stabilization Mechanism in Ultra-Stable Fourier Domain Mode-Locked (FDML) Lasers

Abstract:Understanding the dynamics of Fourier domain mode-locked (FDML) lasers is crucial for determining physical coherence limits, and for finding new superior methods for experimental realization. In addition, the rich interplay of linear and nonlinear effects in a laser ring system is of great theoretical interest. Here we investigate the dynamics of a highly dispersion-compensated setup, where over a bandwidth of more than 100 nm, a highly coherent output with nearly shot-noise-limited intensity fluctuations was experimentally demonstrated. This output is called the sweet-spot. We show by numerical simulation that a finite amount of residual dispersion in the fiber delay cavity of FDML lasers can be compensated by the group delay dispersion in the swept bandpass filter, such that the intensity trace exhibits no dips or high-frequency distortions, which are the main source of noise in the laser. In the same way, a small detuning from the ideal sweep filter frequency can be tolerated. Furthermore, we find that the filter's group delay dispersion improves the coherence properties of the laser, and acts as a self-stabilizing element in the cavity. Our theoretical model is validated against experimental data, showing that all relevant physical effects for the sweet-spot operating regime are included.

Abstract:Passive ultrafast photoelectric devices based on the self-focusing effect have been deeply studied in ultrashort pulse formation, and great progress has been made in solid-state oscillators known as Kerr-lens mode-locking (KLM). The intensity-dependent change of refractive index and the 1-2 fs electronic response time of materials are the basics of KLM. Recently, the advantages of fiber lasers such as compact structure, outstanding environmental stability, excellent heat dissipation potential, and low cost have stimulated great interest among researchers to explore stable and reliable fiber lasers. Based on the feasibility of KML in fiber lasers that have been reported, we demonstrate a high-stable self-mode-locking Er-doped fiber laser in this work. Diverse stable self-mode-locking pulses phenomena can be obtained through adjusting the polarization state of the cavity, including the output pulses with a fundamental frequency of 3.93 MHz, dark-bright soliton pulses, the 3rd harmonic operation, the 81st harmonic operation with the repetition rate of 318.4 MHz and the signal-to-noise ratio of 80 dB, and dual-wavelength output.

Abstract:Harnessing complexity in laser light The development of lasers and the quality of the output light has been crucially dependent on understanding and being able to control the process occurring within the laser-generating cavity. In a real laser cavity, there are both longitudinal and transverse modes; for the highest-quality lasers, reducing the effects of the latter has been standard practice. However, using a graded index fiber cavity, Wright et al. demonstrate that the longitudinal and transverse modes can be locked to provide an output of complex coherent light. Harnessing, rather than filtering out, the transverse modes could produce a valuable and flexible light source applicable across a broad range of disciplines. Science , this issue p. 94

Abstract:Nowadays, mode-locked fiber laser has been extensively applied in various fields such as communication, biomedical, nuclear physics and material processing. By controlling the parameters of cavity elements, people can realize the output of ultrafast pulse with different states. Utilizing the traditional numerical method, the influence of different cavity parameters on the pulses can be computed accurately, which provides the simulation basis for the fabrication of mode-locked fiber lasers. However, with the development of the practical application demand, the performance requirements of the mode-locked pulse are also increasing. The traditional numerical methods have shown some defects in the calculation speed and analysis ability at this time. To improve the shortcomings of the existing numerical methods, in this work, we propose using the machine learning method to analyze the mode-locked pulse convergence of the nonlinear loop mirror (NOLM) fiber mode-locked laser and calculated its pulse information. Firstly, the mapping between cavity parameters and convergence region is established by the support vector machine (SVM) model, and utilizing it, the influence of different cavity pa-rameters on mode-locking is investigated. Then, we train two artificial neural networks (ANN) for calculating the pulse shape and spectral shape in the mode-locked state and find out the cavity parameters under which. the spectral shape approximates to a parabola based on genetic algorithm and the ability of ANN in rapid computing. Finally, we construct the laser cavity according to the numerical result and obtain the mode-locked pulse with a parabolic shape spectrum. The authors believe that the model presented in this work will show widely application prospects in the numerical calculation of fiber lasers.
