Abstract:Streamflow forecasts are traditionally effective in mitigating water scarcity and flood defense. This study developed an artificial intelligence (AI)-based management methodology that integrated multi-step streamflow forecasts and multi-objective reservoir operation optimization for water resource allocation. Following the methodology, we aimed to assess forecast quality and forecast-informed reservoir operation performance together due to the influence of inflow forecast uncertainty. Varying combinations of climate and hydrological variables were input into three AI-based models, namely a long short-term memory (LSTM), a gated recurrent unit (GRU), and a least-squares support vector machine (LSSVM), to forecast short-term streamflow. Based on three deterministic forecasts, the stochastic inflow scenarios were further developed using Bayesian model averaging (BMA) for quantifying uncertainty. The forecasting scheme was further coupled with a multi-reservoir optimization model, and the multi-objective programming was solved using the parameterized multi-objective robust decision-making (MORDM) approach. The AI-based management framework was applied and demonstrated over a multi-reservoir system (25 reservoirs) in the Zhoushan Islands, China. Three main conclusions were drawn from this study: (1) GRU and LSTM performed equally well on streamflow forecasts, and GRU might be the preferred method over LSTM, given that it had simpler structures and less modeling time; (2) higher forecast performance could lead to improved reservoir operation, while uncertain forecasts were more valuable than deterministic forecasts, regarding two performance metrics, i.e., water supply reliability and operating costs; (3) the relationship between the forecast horizon and reservoir operation was complex and depended on the operating configurations (forecast quality and uncertainty) and performance measures. This study reinforces the potential of an AI-based stochastic streamflow forecasting scheme to seek robust strategies under uncertainty.
Assessing Different Roles of Baseflow and Surface Runoff for Long-Term Streamflow Forecasting in Southeastern China

Abstract:Accurate long-term streamflow forecast is essential to alleviate and solve the water security problems related to flood and drought disaster warnings. In this study, a new strategy for forecasting monthly streamflow is proposed and four scenarios are designed for the evaluation of different roles of baseflow and surface runoff on performances of long-term streamflow forecasting. The developed models are evaluated at multiple streamflow sites located in the Zhejiang Province of China. The results show that artificial intelligence (AI)-based models with two predictor variables (i.e. baseflow and surface runoff) performed better than that with a single predictor (streamflow) for all the months in a year, and the prediction accuracy of annual peak and monthly streamflow values is improved. Based on the comprehensive evaluations of all the models, the baseflow and surface runoff values are recommended as inputs to AI-based models for an improved prediction accuracy of streamflows.
Attribution of Hydrologic Forecast Uncertainty Within Scalable Forecast Windows

Abstract:Hindcasts based on the extended streamflow prediction (ESP) approach are carried out in a typical rainfall-dominated basin in China, aiming to examine the roles of initial conditions (IC), future atmospheric forcing (FC) and hydrologic model uncertainty (MU) in streamflow forecast skill. The combined effects of IC and FC are explored within the framework of a forecast window. By implementing virtual numerical simulations without the consideration of MU, it is found that the dominance of IC can last up to 90 days in the dry season, while its impact gives way to FC for lead times exceeding 30 days in the wet season. The combined effects of IC and FC on the forecast skill are further investigated by proposing a dimensionless parameter (β) that represents the ratio of the total amount of initial water storage and the incoming rainfall. The forecast skill increases exponentially with β, and varies greatly in different forecast windows. Moreover, the influence of MU on forecast skill is examined by focusing on the uncertainty of model parameters. Two different hydrologic model calibration strategies are carried out. The results indicate that the uncertainty of model parameters exhibits a more significant influence on the forecast skill in the dry season than in the wet season. The ESP approach is more skillful in monthly streamflow forecast during the transition period from wet to dry than otherwise. For the transition period from dry to wet, the low skill of the forecasts could be attributed to the combined effects of IC and FC, but less to the biases in the hydrologic model parameters. For the forecasts in the dry season, the skill of the ESP approach is heavily dependent on the strategy of the model calibration.
Differing roles of base and fast flow in ensemble seasonal streamflow forecasting: An experimental investigation

Abstract:<p>Seasonal streamflow forecasting, which is important for water resources management, is generally a challenging task in hydrology. This paper focuses on the consideration of base and fast flow for the forecasting of seasonal streamflow. Taking the three tributaries of the Pearl River in South China as case study, five forecasting experiments, which forecast the average daily flow in the three-month period by using the average daily flow in the antecedent month, are devised to elucidate the different roles of base, fast, and total flow. The recursive digital filter (RDF) model is employed for the separation of base flow from fast flow; the Bayesian joint probability (BJP) model is applied to generate ensemble forecasts under cross validation; and the Schaake shuffle is used to establish temporal structure to link ensemble members when adding up forecasts of base flow and fast flow. Forecasts in the different experiments are evaluated in terms of bias, reliability, and skill, and the relationship between correlation coefficient and forecast skill is illustrated. The results show that unbiased and reliable seasonal forecasts are generally obtained in the experiments. Correlation coefficients of base flow are overall higher than those of total flow while correlation coefficients of fast flow are lower. Forecast skill tends to increase with correlation coefficient. Meanwhile, fast flow can lead to extremely large total flow in the antecedent month, which can substantially enlarge the forecasts and diminish the forecast skill when the corresponding observation is not as large. By contrast, base flow tends to always contribute to forecast skill. The separation of base flow from fast flow, which accounts for the different dynamical processes of fast and base flow, can reduce the impact of fast flow and improve the forecast skill of total flow.</p>

Abstract:The non-stationary, complex, and non-linear characteristics of streamflow time series have a significant impact on the simulation results of the conventional hydrological forecasting models. To improve the performances, this paper develops an enhanced machine learning model for streamflow time series forecasting, where the twin support vector regression (TSVR) is combined with singular spectrum analysis (SSA) and grey wolf optimizer (GWO). Specially, the SSA method is set as the data preprocessing tool for pattern identification; the TSVR model is set as the basic forecasting module for each pattern and the GWO method is used as the optimizer to select feasible parameter combination. Multi-step-ahead streamflow forecasting tasks are used to examine the feasibility and predictability of the proposed model. The results indicate that the proposed model can yield superior results compared with the traditional forecasting models. Thus, a robust and reliable tool is provided for streamflow time series forecasting under uncertainty.

Abstract:Abstract. A popular way to forecast streamflow is to use bias-corrected meteorological forecasts to drive a calibrated hydrological model, but these hydrometeorological approaches suffer from deficiencies over small catchments due to uncertainty in meteorological forecasts and errors from hydrological models, especially over catchments that are regulated by dams and reservoirs. For a cascade reservoir catchment, the discharge from the upstream reservoir contributes to an important part of the streamflow over the downstream areas, which makes it tremendously hard to explore the added value of meteorological forecasts. Here, we integrate meteorological forecasts, land surface hydrological model simulations and machine learning to forecast hourly streamflow over the Yantan catchment, where the streamflow is influenced by both the upstream reservoir water release and the rainfall–runoff processes within the catchment. Evaluation of the hourly streamflow hindcasts during the rainy seasons of 2013–2017 shows that the hydrometeorological ensemble forecast approach reduces probabilistic and deterministic forecast errors by 6 % compared with the traditional ensemble streamflow prediction (ESP) approach during the first 7 d. The deterministic forecast error can be further reduced by 6 % in the first 72 h when combining the hydrometeorological forecasts with the long short-term memory (LSTM) deep learning method. However, the forecast skill for LSTM using only historical observations drops sharply after the first 24 h. This study implies the potential of improving flood forecasts over a cascade reservoir catchment by integrating meteorological forecasts, hydrological modeling and machine learning.

Abstract:Hydrological ensemble forecasting is crucial for flood forecasting. However, the centralized architecture of hydrological ensemble forecasting systems requires time- and labour-intensive downloads and the installation of executable models and methods. This usage pattern impedes the reusability of forecasting models and techniques. To address these limitations, we propose an open online simulation strategy with three components: model sharing and integration, data sharing and adaptation, and parameter optimization and recommendation. The model sharing and integration method helps researchers publish forecasting models as web services for online simulation and integration. A reusable data sharing and adaptation method is established for managing and processing data to meet model requirements. In addition, the optimization and recommendation methods are intended to assist researchers in optimizing and recommending model parameters online based on the characteristics of different research regions. Finally, a prototype system and case study are constructed to verify the strategy's feasibility and capability.

Abstract:Accurate, reliable, and stable streamflow forecasts are essential for risk assessment and decision making in water resources management. Owing to the limited value of deterministic forecasting, probabilistic forecasting incorporating probability and confidence intervals is achieved by optimizing the predictors and forecast equation while identifying forecast error features. The combination of deterministic forecasts and error identification can facilitate water resources management. This study improved the traditional forecast model's inputs selection, structure designation, and error parameters calibration to propose a long-term probabilistic streamflow forecast model with hierarchical optimization of the predictors, forecast equation, and errors characteristics. The model develops information entropy theory to screen the driving predictor set, the long short-term memory (LSTM) model to conduct deterministic forecasts, and the generalized autoregressive conditional heteroskedasticity (GARCH) model to identify time-varying errors. The proposed model, used in some case studies to forecast the monthly streamflow of two lakes, Hongze and Luoma lakes in China, was evaluated using the multidimensional index method considering "accuracy-reliability-stability" performance. The results revealed the following: (1) Predictor screening based on information entropy investigates the statistical characteristics of predictors, thereby improving the reliability of streamflow forecasts. (2) The LSTM model exploits the response between the driving predictors and streamflow, whereas GARCH model identifies the time-varying features of forecast errors effectively, which reduces the probability of forecast failure and increases the accuracy and stability of probabilistic forecasts. (3) Under current meteorological observation conditions and forecasting capability, the proposed forecasts can extend the maximum forecast lead time from 1 month to 3 months. (4) The proposed model improves the accuracy (root mean square error: 6.7%-34.8%), reliability (Brier score: 15.3%-27.9%), and stability (mistaken distance: 36.4-52.6%) in comparison with the benchmark of the two case studies, indicating that "inputs-structure-parameters" hierarchical optimization provides effective forecast information for water resources management.

Abstract:Streamflow simulation is of great importance for water engineering design and water resource management. Most existing models simulate streamflow by establishing a quantitative relationship among climate, human activities, and streamflow and assuming the relationship is stationary in the long term. However, in a changing environment, this relationship may vary over time, resulting in the poor performance of many existing streamflow simulation models. In this study, inspired by data stream mining, adapting the gradient-boosted regression tree (XGBoost) to work in an online setting, a new statistically based model, called an online gradient-boosted regression tree (online XGBoost), is proposed to simulate streamflow dynamically in a changing environment. Here, the data of streamflow, climatic variables, and human activities are regarded as a data stream and the change in their relationships is treated as concept drift. The proposed model has two attractive properties. First, it makes it possible to capture the changed relationship between streamflow and its impact factors with the concept of a drift detection algorithm. Second, it can be used to simulate streamflow dynamically by updating models based on the concept drift detection results. Taking the Qingliu River catchment as a case study, the results show that the proposed method achieved good performance on monthly streamflow simulations during 1989 and 2010 with a Nash-Sutcliffe model efficiency coefficient (NSE) of 0.73. Furthermore, it outperformed comparable methods, including four statistically based methods (online support vector regression, online regression tree, online random forest regression, and online boosting tree regression) and four lumped parameter hydrological models (SimHyd, Sacramento, soil moisture accounting and routing, and Tank). The proposed model provides a useful tool for streamflow simulation in a changing environment. Findings will help water resource managers adapt to climate change.

Abstract:Stochastic nature of streamflow poses significant challenges in attaining a reliable forecasting model. In general, variational mode decomposition (VMD) can improve the forecast performance but easily expose the sub-signals to boundary effect. Furthermore, one model is not able to adapt all properties of different sub-series. Accordingly, we have two aims in this study. One is to propose an adaptive weight combined forecasting model to improve the middle and long-term streamflow forecast skill. It adapts the boundary effect in such a way that its inputs come from decomposition during calibration sets, and outputs are extracted from decomposition during the entire series. The other one is to link system performance improvement, i.e., the forecast skill, to the forecast value to address the gap in methodologies appropriate for data-limited locations (only hydrological time series collected). Four artificial intelligence-based models coupled with adaptive appendant and parameter optimization are developed as hybrid adaptive (HA) for forecasting each sub-signal decomposed by VMD in the proposed forecast model. The multi-objective grey wolf optimization (MOGWO) algorithm is then employed to combine individual forecasts based on performance-based weighting strategies and provide the Pareto-optimal ensemble forecasts. The proposed model is applied to forecast streamflow 1 to 6 months ahead of two stations in the Yellow River, China, and the results show that the ensemble forecasts can increase the values of Nash-Sutcliffe efficiency coefficient by 0.10 ~ 7.96% and reducing the values of root mean squared error by 1.08 ~ 32.11% compared to the HA model. The relationship between the forecast skill and its value can be strongly affected by decision-makers priorities, but the relative improvement in hydropower generation obtained by the compromised forecasts going from 0.02% to 3.39% indicates that improved forecasts are potentially valuable for informing strategic decisions.

Abstract:Streamflow, as a natural phenomenon, is continuous in time and so are the meteorological variables which influence its variability. In practice, it can be of interest to forecast the whole flow curve instead of points (daily or hourly). To this end, this paper introduces the functional linear models and adapts it to hydrological forecasting. More precisely, functional linear models are regression models based on curves instead of single values. They allow to consider the whole process instead of a limited number of time points or features. We apply these models to analyse the flow volume and the whole streamflow curve during a given period by using precipitations curves. The functional model is shown to lead to encouraging results. The potential of functional linear models to detect special features that would have been hard to see otherwise is pointed out. The functional model is also compared to the artificial neural network approach and the advantages and disadvantages of both models are discussed. Finally, future research directions involving the functional model in hydrology are presented.
A Forecast-Skill-Based Dynamic Pre-Storm Level Control for Reservoir Flood-Control Operation

Abstract:The design and operation of reservoirs based on conventional flood-limited water levels (FLWL) implicitly adopts the assumption of hydrological stationarity. As such, historical-record-based FLWL may not be the best choice for flood-control operations due to the inherent non-stationarity of rainfall inputs. With maturing flood forecasts, this study focuses on establishing linkage between FLWL and skill of forecast, thus developing a “dynamic pre-storm level” approach for reservoir flood-control operations. The approach utilizes forecast flood magnitude, forecast skill and exceedance probability of forecast error to determine the pre-storm reservoir storage for each flood event. The exceedance probability of forecast error for each incoming flood is used as the reservoir flood control standard instead of the probability of a static return interval flood. This approach is demonstrated in a hypothetical situation in the Three Gorges Reservoir in China. The results show that under zero-forecast-skill conditions, the proposed dynamic pre-storm level matches well with the Three Gorges Reservoir-designed FLWL; and, as the forecast accuracy/skill increase, the proposed approach can make better use of the increased forecast accuracy, thereby maximizing floodwater utilization and reservoir storage. In this way, coupling the new approach with FLWL allows for more efficient and economic day-to-day reservoir operations without adding any flood risk. This study validates the usefulness of dynamic water level control during flood season, considering the improvement of flood forecast accuracy.

Abstract:With the goal of forecasting streamflow time series with sufficient lead time, we evaluate the efficiency and accuracy of data-based models ranging from relatively simple to complex. Based on this, we systematically explain the model construction and selection process according to lead time, type and amount of data, and optimization method. This analysis involved optimizing the inputs and hyperparameters of four unique data-driven models: Autoregressive Integrated Moving Average (ARIMA), Artificial Neural Network (ANN), Long Short-Term Memory (LSTM), and Transformer (TRANS), which were applied to the Soyang watershed, South Korea. The type and amount of model inputs are determined through a fine-tuning process that samples based on a correlation threshold, correlation to predictand, and autocorrelation to historical data and evaluates the simulated objective function. Hyperparameters are simultaneously optimized using three conventional optimization methods: Bayesian optimization (BO), particle swarm optimization (PSO), and gray wolf optimization (GWO). The experimental results provide insight into the role of input predictors, data preparations (e.g., wavelet transform), hyperparameter optimization, and model structures. From this, we can provide guidelines for model selection. Relatively simple models can be used when the dataset is small or there are few input variables, when only the near future is predicted, or when the selection of optimization methods is limited. However, a more complex model should be selected if the type and amount of data are sufficient, various optimization methods can be applied, or it is necessary to secure more lead time. More parameters, more complex model structures, and more training materials make this possible.

Multi-Variables-Driven Model Based on Random Forest and Gaussian Process Regression for Monthly Streamflow Forecasting

Abstract:Due to the inherent non-stationary and nonlinear characteristics of original streamflow and the complicated relationship between multi-scale predictors and streamflow, accurate and reliable monthly streamflow forecasting is quite difficult. In this paper, a multi-scale-variables-driven streamflow forecasting (MVDSF) framework was proposed to improve the runoff forecasting accuracy and provide more information for decision-making. This framework was realized by integrating random forest (RF) and Gaussian process regression (GPR) with multi-scale variables (hydrometeorological and climate predictors) as inputs and is referred to as RF-GPR-MV. To validate the effectiveness and superiority of the RF-GPR-MV model, it was implemented for multi-step-ahead monthly streamflow forecasts with horizons of 1 to 12 months for two key hydrological stations in the Jinsha River basin, Southwest China. Other MVDSF models based on the Pearson correlation coefficient (PCC) and GPR with/without multi-scale variables or the PCC and a backpropagation neural network (BP) or general regression neural network (GRNN), with only previous streamflow and precipitation, namely, PCC-GPR-MV, PCC-GPR-QP, PCC-BP-QP, and PCC-GRNN-QP, respectively, were selected as benchmarks. Experimental results indicated that the proposed model was superior to the other benchmark models in terms of the Nash–Sutcliffe efficiency (NSE) for almost all forecasting scenarios, especially for forecasting with longer lead times. Additionally, the results also confirmed that the addition of large-scale climate and circulation factors was beneficial for promoting the streamflow forecasting ability, with an average contribution rate of about 15%. The RF in the MVDSF framework improved the forecasting performance, with an average contribution rate of about 25%. This improvement was more pronounced when the lead time exceeded 3 months. Moreover, the proposed model could also provide prediction intervals (PIs) to characterize forecast uncertainty, as supplementary information to further help decision makers in relevant departments to avoid risks in water resources management.

Abstract:Skillful streamflow forecasts can inform decisions in various areas of water policy and management. We integrate numerical weather prediction ensembles, distributed hydrological models, and machine learning to generate ensemble streamflow forecasts at medium-range lead times (1–7 days). We demonstrate a case study for machine learning applications in postprocessing ensemble streamflow forecasts in the Upper Susquehanna River basin in the eastern United States. Our results show that the machine learning postprocessor can improve streamflow forecasts relative to low-complexity forecasts (e.g., climatological and temporal persistence) as well as standalone hydrometeorological modeling and neural network. The relative gain in forecast skill from postprocessor is generally higher at medium-range timescales compared to shorter lead times; high flows compared to low–moderate flows, and the warm season compared to the cool ones. Overall, our results highlight the benefits of machine learning in many aspects for improving both the skill and reliability of streamflow forecasts.

Abstract:This paper aims to introduce an artificial intelligence approach to enhance short-term daily streamflow forecasts through the integration of machine learning (ML) techniques with meta -heuristic (MH) algorithms. To maximize performance, a comprehensive analysis involving the autocorrelation and partial autocorrelation functions of the observed streamflow was conducted to derive ten distinct input combinations, from which the most suitable set was selected for investigation. Subsequently, six distinct ML methods, namely, decision trees , support vector regression , long short-term memory, gated recurrent unit, multi-layer perceptron , and radial basis function (as the optimal input combination), were leveraged to predict one-day-ahead streamflow. The most promising outcomes from these six explored methods were synergistically amalgamated to enhance predictive precision. This amalgamation was then optimized by utilizing parameter values hyper-tuned by four different MH algorithms. The algorithms included the shuffled frog leaping algorithm, particle swarm optimization , ant colony optimization (ACO), and gray wolf optimization (GWO). In culmination, a case study centered around the "Wick" river in the UK was conducted to rigorously evaluate the performance of the proposed method, utilizing a range of statistical evaluation indices. The results underscored the efficacy of the proposed combined method in substantially refining streamflow predictions, exhibiting an impressive level of accuracy. Additionally, the outcomes emphasized that ACO and GWO stand out as the optimal algorithms for calibrating the parameters of the amalgamated model. For instance, the R 2 values attained by the combined models optimized through the ACO and GWO algorithms were 0.69422 and 0.69444, respectively. These values notably surpass those observed in the initial models, substantiating the superiority of the applied optimization approaches.

Abstract:<p>Long-term streamflow forecasting for a multisite river basin system can experience oscillation of spatio-temporal dependent forecast errors. Characterizing the dependent information and conducting spatio-temporal dependent forecast error correction can reduce the total uncertainty in real-time forecasting. On the basis of a single-site martingale model of forecast evolution (MMFE), which can simulate forecast uncertainty evolution over the temporal scale, this study developed a dynamic long-term streamflow probabilistic forecasting model that addresses spatio-temporal dependent error correction for a multisite system. Error characteristics and hybrid spatio-temporal forecast improvements with complex dependencies are captured by Copula function, which describes the systemwide evolution of forecast uncertainty. The proposed model was verified by forecasting the streamflow of the Hongze Lake–Luoma Lake system in China. The results revealed the following. 1) The spatio-temporal dependent error correction based on MMFE can refine the spatio-temporal dimension hybrid error information, which is helpful in improving forecast accuracy. 2) As the spatio-temporal dependence of forecast uncertainty is described using a Copula function, selection of the marginal distribution and connection function is flexible through combining statistical and informational characteristics of the errors, which is helpful in improving the fittedness of complex system error simulation. 3) Compared with the benchmark forecast model without correction, the proposed model greatly decreased forecast uncertainty by reducing the standard deviation of the errors, continuous ranked probability score (CRPS), and Brier score (BS) by nearly 40%, 11.4%, and 34.6%, respectively, and further reduce the CRPS by 2.1% on average (highest value: 3.7%) and reduce the BS by 1.2% on average (highest value: 2.0%) in comparison with only temporal correction. The results demonstrate that the proposed model improves the accuracy and reliability of probabilistic streamflow forecasting for complex water resource systems by reducing uncertainty.</p>

Abstract:Study region The Yarlung Zangbo River (YZR) basin on the Tibetan Plateau, China Study focus Due to global climate change, the risk of drought disaster is increasing. Seasonal hydrological forecast can be beneficial for drought early warning and help reduce risks in water resources and drought management. However, the computational burden of distributed hydrological models remains a limitation for their wide use in seasonal streamflow forecast. This study designs a seasonal streamflow forecast framework based on the surrogate model (SM) for VIC. Both the impacts of pre-processing and post-processing on the seasonal streamflow forecast, and the accuracy, reliability and efficiency of the forecast framework based on SM, are carefully evaluated in the YZR basin, China. New hydrological insights for the region The results show that the VIC model forced by CFSv2 has a good predictability and reliability in seasonal streamflow forecast in the YZR basin. Both pre-processing and post-processing can improve streamflow forecast accuracy, while post-processing also improves the forecast reliability more significantly. The SM-simulated streamflow is identical with that of VIC, with NSE larger than 0.95 and Pbias smaller than 5% at Nuxia station, in the YZR basin. The proposed SM-based seasonal streamflow forecast framework has been proven to be a good alternative for the VIC-based framework, with similar forecast accuracy and reliability, and higher computational efficiency, reducing up to 97% computation time.

Abstract:Stream-flow forecasting for small rivers has always been of great importance, yet comparatively challenging due to the special features of rivers with smaller volume. Artificial Intelligence (AI) methods have been employed in this area for long, but improvement of forecast quality is still on the way. In this paper, we tried to provide a new method to do the forecast using the Long-Short Term Memory (LSTM) deep learning model, which aims in the field of time-series data. Utilizing LSTM, we collected the stream flow data from one hydrologic station in Tunxi, China, and precipitation data from 11 rainfall stations around to forecast the stream flow data from that hydrologic station 6 hours in the future. We evaluated the prediction results using three criteria: root mean square error (RMSE), mean absolute error (MAE), and coefficient of determination (R^2). By comparing LSTM's prediction with predictions of Support Vector Regression (SVR) and Multilayer Perceptions (MLP) models, we showed that LSTM has better performance, achieving RMSE of 82.007, MAE of 27.752, and R^2 of 0.970. We also did extended experiments on LSTM model, discussing influence factors of its performance.

Abstract:In order to overcome the shortcoming of the solution may be trapped into the local minimization in the traditional TSK (Takagi-Sugeno-Kang) fuzzy inference training, this paper attempts to consider the TSK fuzzy system modeling approach based on the visual system principle and the Weber law. This approach not only utilizes the strong capability of identifying objects of human eyes, but also considers the distribution structure of the training data set in parameter regulation. In order to overcome the shortcoming of it adopting the gradient learning algorithm with slow convergence rate, a novel visual TSK fuzzy system model based on evolutional learning is proposed by introducing the particle swarm optimization algorithm. The main advantage of this method lies in its very good optimization, very strong noise immunity and very good interpretability. The new method is applied to long-term hydrological forecasting examples. The simulation results show that the method is feasibile and effective, the new method not only inherits the advantages of traditional visual TSK fuzzy models but also has the better global convergence and accuracy than the traditional model.
