Abstract:A water demand forecasting model based on artifical neural networks (ANN) was proposed. To overcome the slow convergence rate of the classic BP method. The new learnimg algirithm introduced a variable-schedule method with adaptive step and momentum in training of the feedforward neural metwdork. As many factors influencing water demand are taken into accoumt, the forecasting model proposed is capable of elementary system delision-making. A case study shows that the forecasting model and its corresponding method has good precision and accuracy. In order to improve the learning efficiency of multi-layer feedforward neural network, a variable-schedule method was introduced to train the weights of neural network. According to the training errors, the learning coefficients and the momentum factors were self-adaptively adjusted. Applying this method to forecast urban water demand, a forecasting model of nonlinear artificial neural network was established, which included the influences of many factors to urban water demand, such as repeated utilization ratio of industrial water, population, economic development and so on. The proposed forecastion model has systematic decision-making function. The application examples in Hangzhou city show that the forecasting model and its corresponding calculating method has higher forecasting precision and accuracy.
A two-stage surrogate model based on ANN and AdaBoost for multi-objective parameter optimization of the Variable Infiltration Capacity model

Abstract:Distributed hydrologic models have been widely used for its functional diversity and rationality in theory. However, calibration of distributed models is computationally expensive with a large number of model runs, even if an efficient multi-objective algorithm is employed. To alleviate the burden of computation, we develop a two-stage surrogate model by coupling backpropagation neural network with AdaBoost to calibrate the parameters of the Variable Infiltration Capacity (VIC) model. The first stage model selects the parameter sets with simulated outputs in the crucial range and the second stage model estimates the values of outputs accurately with the parameter sets picked out by the first stage model. The developed surrogate model is tested in three different river basins in China, namely the Lanjiang River basin (LJR), the Xiangjiang River basin (XJR) and the Upper Brahmaputra River basin (UBR). With sufficient samples generated by ε-NSGA II, the surrogate model performs very well with a low error rate of classification (ER) and root mean square error (RMSE). The streamflow simulated with the surrogate model is nearly the same as that from the original VIC model, indicating that the surrogate model does gain a remarkable speedup compared with the original VIC model.
Support Vector Machine―an Alternative to Artificial Neuron Network for Water Quality Forecasting in an Agricultural Nonpoint Source Polluted River?

Abstract:Water quality forecasting in agricultural drainage river basins is difficult because of the complicated nonpoint source (NPS) pollution transport processes and river self-purification processes involved in highly nonlinear problems. Artificial neural network (ANN) and support vector model (SVM) were developed to predict total nitrogen (TN) and total phosphorus (TP) concentrations for any location of the river polluted by agricultural NPS pollution in eastern China. River flow, water temperature, flow travel time, rainfall, dissolved oxygen, and upstream TN or TP concentrations were selected as initial inputs of the two models. Monthly, bimonthly, and trimonthly datasets were selected to train the two models, respectively, and the same monthly dataset which had not been used for training was chosen to test the models in order to compare their generalization performance. Trial and error analysis and genetic algorisms (GA) were employed to optimize the parameters of ANN and SVM models, respectively. The results indicated that the proposed SVM models performed better generalization ability due to avoiding the occurrence of overtraining and optimizing fewer parameters based on structural risk minimization (SRM) principle. Furthermore, both TN and TP SVM models trained by trimonthly datasets achieved greater forecasting accuracy than corresponding ANN models. Thus, SVM models will be a powerful alternative method because it is an efficient and economic tool to accurately predict water quality with low risk. The sensitivity analyses of two models indicated that decreasing upstream input concentrations during the dry season and NPS emission along the reach during average or flood season should be an effective way to improve Changle River water quality. If the necessary water quality and hydrology data and even trimonthly data are available, the SVM methodology developed here can easily be applied to other NPS-polluted rivers.

Abstract:Accurate forecasting of annual runoff time series is of great significance for water resources planning and management. However, considering that the number of forecasting factors is numerous, a single forecasting model has certain limitations and a runoff time series consists of complex nonlinear and nonstationary characteristics, which make the runoff forecasting difficult. Aimed at improving the prediction accuracy of annual runoff time series, the principal components analysis (PCA) method is adopted to reduce the complexity of forecasting factors, and a modified coupling forecasting model based on multiple linear regression (MLR), back propagation neural network (BPNN), Elman neural network (ENN), and particle swarm optimization-support vector machine for regression (PSO-SVR) is proposed and applied in the Dongbei Hydrological Station in the Ganjiang River Basin. Firstly, from two conventional factors (i.e., rainfall, runoff) and 130 atmospheric circulation indexes (i.e., 88 atmospheric circulation indexes, 26 sea temperature indexes, 16 other indexes), principal components generated by linear mapping are screened as forecasting factors. Then, based on above forecasting factors, four forecasting models including MLR, BPNN, ENN, and PSO-SVR are developed to predict annual runoff time series. Subsequently, a coupling model composed of BPNN, ENN, and PSO-SVR is constructed by means of a multi-model information fusion taking three hydrological years (i.e., wet year, normal year, dry year) into consideration. Finally, according to residual error correction, a modified coupling forecasting model is introduced so as to further improve the accuracy of the predicted annual runoff time series in the verification period.

Abstract:In recent decades, the daily runoff forecasting based on artificial Neural Network (ANN) models has become quite important to deliver sustainable use and effective planning and management of water resources. The performance of the existent ANN models for 1 day in advance forecasting are frequently reported. However, the mid-term forecasting by ANN is scarce in the literature. In this study, a feed forward network trained with a back-propagation learning algorithm (BP-ANN) is used to construct a mid-short-term daily runoff forecasting system. ANN models having various input variables were constructed and the best structure was investigated. Moreover, the performance of ANN models and multiple process-based rainfall-runoff models, including Xinanjiang, ESSI, SWAT and XXT, is compared. Baohe River basin, located in central China, is chosen as a case study area. The results show that in general the performance of ANN models decrease as the lead time increase when the lead time is less than 11 days; while it varies slightly with lead time when the lead time is larger than 11 days. The ANN model with an appropriate combination of stream flow, precipitation as input variables performs much better than all the process-based rainfall-runoff models in terms of Nash-Sutcliffe efficiency for mid-short-term daily runoff forecasting.

Abstract:In this paper, a novel ANN flood forecasting model is proposed. The ANN model is combined with traditional hydrological concepts and methods, taking the initial Antecedent Precipitation Index (API), rainfall, upstream inflow and initial flow at the forecast river section as input of model, and flood flow forecast of the next time steps as output of the model. The distributed rainfall is realized as the input of the model. The simulation is processed by dividing the watershed into several rainfall-runoff processing units. Two hidden layers are used in the ANN, and the topology of ANN is optimized by connecting the hidden layer neurons only with the input which has physical conceptual causes. The topological structure of the proposed ANN model and its information transmission process are more consistent with the physical conception of rainfall-runoff, and the weight parameters of the model are reduced. The arithmetic moving-average algorithm is added to the output of the model to simulate the pondage action of the watershed. Satisfactory results have been achieved in the Mozitan and Xianghongdian reservoirs in the upper reaches of Pi river in Huaihe Basin, and the Fengman reservoir in the upper reach of Second Songhua river in Songhua basin in China.

Abstract:The rainfall–runoff relationship is not only nonlinear and complex but also difficult to model. Artificial neural network (ANN), as a data-driven technique, has gained significant attention in recent years and has been shown to be an efficient alternative to traditional methods for hydrological modeling. However, for different input combinations, ANN models can yield different results. Therefore, input variables and ANN types need to be carefully considered, when using an ANN model for stream flow forecasting. This study proposes the copula-entropy (CE) theory to identify the inputs of an ANN model. The CE theory permits to calculate mutual information (MI) and partial MI directly which avoids calculating the marginal and joint probability distributions. Three different ANN models, namely multi-layer feed (MLF) forward networks, radial basis function networks and general regression neural network, were applied to predict stream flow of Jinsha River, China. Results showed that the inputs selected by the CE method were better than those by the traditional linear correlation analysis, and the MLF ANN model with the inputs selected by CE method obtained the best predicted results for the Jinsha River at Pingshan gauging station.

Abstract:Accurate long-term runoff forecasting is crucial for managing and allocating water resources. Due to the complexity and variability of natural runoff, the most difficult problems currently faced by long-term runoff forecasting are the difficulty of model construction, poor prediction accuracy, and time intensive forecasting processes. Therefore, this study proposes a hybrid long-term runoff forecasting framework that uses the antecedent inflow and specific meteorological factors as the inputs, is modeled by ensemble empirical mode decomposition (EEMD) coupled with an artificial neural network (ANN), and computed by a parallel algorithm. First, the framework can transform monthly inflow and meteorological series into stationary signals via EEMD to more comprehensively explore the relationships of the input factors through the ANN. Second, the selected meteorological factors that are closely related to inflow formation can be filtered out by the single correlation coefficient method, which contributes to reducing coupling between input factors, and increases the accuracy of the prediction models. Finally, a multicore parallel algorithm that is easily accessed everywhere and that fully utilizes multiple calculation resources while flexibly contending with various optimization requirements will improve forecasting efficiency. The Xiaowan Hydropower Station (XW) is selected as the study area, and the final results of the study show that (1) the addition of targeted meteorological factors does indeed greatly enhance the performance of the prediction models; (2) the five criteria for evaluating the prediction accuracy show that the EEMD-ANN model is far superior to the prediction performance from the ordinary ANN model when run under the same input conditions; and (3) the optimization time of the 32-core model can be reduced by as much as 25 times, which significantly saves time during the forecast process.

Prediction of Soil-Water Characteristic Curve Using Artificial Neural Network Approach

Abstract:In pavement ME design, the soil-water characteristic curve (SWCC) is used to estimate the resilient modulus of unbound material at different saturation conditions based on the enhanced integrated climatic model (EICM). The Fredlund-Xing equation is employed to generate the SWCC and the fitting parameters of the equation are correlated to the soil physical properties using regression models. However, the prediction accuracy of this method needs to be improved. To solve this problem, this study employs an artificial neural network (ANN) approach to improve the prediction accuracy of the SWCC fitting parameters. A new set of SWCC-related soil physical properties are selected to predict the SWCC. A large number of soil datasets collected from the NCHRP 9-23A project are used to develop the ANN models. The developed ANN models of the SWCC fitting parameters are used to predict the suction-water content relationship. The R-2 values were found to be 0.9 and 0.95 for predicting the SWCC curves of plastic and non-plastic soils respectively, which are significantly higher than existing correlation models. The prediction accuracy of the developed ANN models are validated by comparing the measured and predicted matric suction of new soils datasets that are not used to train the ANN models.

Abstract:Accurate and consistent annual runoff prediction in a region is a hot topic in management, optimization, and monitoring of water resources. A novel prediction model (ESMD-SE-WPD-LSTM) is presented in this study. Firstly, extreme-point symmetric mode decomposition (ESMD) is used to produce several intrinsic mode functions (IMF) and a residual (Res) by decomposing the original runoff series. Secondly, sample entropy (SE) method is employed to measure the complexity of each IMF. Thirdly, wavelet packet decomposition (WPD) is adopted to further decompose the IMF with the maximum SE into several appropriate components. Then long short-term memory (LSTM) model, a deep learning algorithm based recurrent approach, is employed to predict all components. Finally, forecasting results of all components are aggregated to generate the final prediction. The proposed model, which is applied to seven annual series from different areas in China, is evaluated based on four evaluation indexes (R, MAE, MAPE and RMSE). Results indicate that ESMD-SE-WPD-LSTM outperforms other benchmark models in terms of four evaluation indexes. Hence the proposed model can provide higher accuracy and consistency for annual runoff prediction, rendering it an efficient instrument for scientific management and planning of water resources.

Abstract:Numerous studies have demonstrated that the combination models can improve the runoff forecast performance compared to individual forecasts. However, some models do not take into account the effects of inappropriate sub-models on the combination models. Based on this, a medium-and long-term runoff integrated forecasting method based on optimal sub-models selection was proposed. Firstly, the sub-models, including linear regression (MLR), BP neural network (BPNN), wavelet neural network (WNN), and support vector regression (SVR), are optimally selected based on the nearness degree. Secondly, RR is used to combine the optimal sub-models to predict runoff. Finally, the Guandi hydropower station is taken as an example to verify the effect of the integrated forecasting model. The results show that SVR, BPNN, and WNN are the optimal sub-models, and RR-3 is the optimal integrated forecasting model composed of the optimal sub-models. In addition, compared with the other two combination models, the RR-3 performs better.

Abstract:Abstract Accurate daily runoff prediction plays an important role in the management and utilization of water resources. In order to improve the accuracy of prediction, this paper proposes a deep neural network (CAGANet) composed of a convolutional layer, an attention mechanism, a gated recurrent unit (GRU) neural network, and an autoregressive (AR) model. Given that the daily runoff sequence is abrupt and unstable, it is difficult for a single model and combined model to obtain high-precision daily runoff predictions directly. Therefore, this paper uses a linear interpolation method to enhance the stability of hydrological data and apply the augmented data to the CAGANet model, the support vector machine (SVM) model, the long short-term memory (LSTM) neural network and the attention-mechanism-based LSTM model (AM-LSTM). The comparison results show that among the four models based on data augmentation, the CAGANet model proposed in this paper has the best prediction accuracy. Its Nash–Sutcliffe efficiency can reach 0.993. Therefore, the CAGANet model based on data augmentation is a feasible daily runoff forecasting scheme.

Abstract:The generation of runoff was affected by several factors.Runoff series always contain information of multiple factors,which make the variation of runoff complex.People usually model the regular pattern of the hydrologic time series by applying a univariate artificial neural network(ANN) model to simulate the variational process.However,it is often unacceptable because of the low prediction precision.We analyze the variation of the hydrologic time series and deseasonalize and detrend it before inputting it for ANN training data.The results show that the ANN that uses processed training data excelled the ANN that uses original data for training data.Meanwhile,we detect the fractal characteristic of the hydrologic time series and estimate the range of invariant scale employing the detrend fluctuation analysis(DFA) method.We choose different numbers of training data and get corresponding ANN models.The results of the experiments indicate that we have more chances to obtain the best ANN model when select a training data with a number with in the scale range.
Integration Of Ann With Topmodel In Daily Stream Flow Forecasting

Abstract:Despite the strength and a increasing interest in application of artificial neural networks (ANNs) to rainfall runoff simulating, the deficiencies associated with traditional applications of ANNs in which the networks essentially function as black box models is obvious. The objective of this work is therefore to enhance the ANN-based rainfall runoff models' ability in the description of hydrological processes such as interception, infiltration, surface runoff, sub-surface runoff and evapotranspiration by integrating it with TOPMODEL, which is a simple physically based rainfall-runoff model and has become increasingly popular and widely used in a great number of applications in recent years. A new integrated model named ANN-TOPMODEL is proposed in this study. Baohe River basin (2413 km(2)), located at the upper stream of the Hanjiang Catchment in Yangtze River Basin, China, is selected as the study area for testing the new model. The results show that the daily stream flows simulated by the new model are in good agreement with the observed ones, while the daily stream flows simulated by TOPMODEL greatly overestimates or underestimates some peak flows both for calibration period and validation period. Further more, the new model resulted in a Nash and Sutcliffe efficiency coefficient value of 0.905 for validation period, which is significantly larger than TOPMODEL. The results demonstrate that the proposed integrated model based on ANN and TOPMODEL is promising in daily stream flow modeling.
Stream Flow Forecasting by Artificial Neural Network and TOPMODEL in Baohe River Basin

Abstract:Black box-based ANN (artificial neural network) models and the process-based model TOPMODEL have been increasingly applied to various water resources system problems in recent years. One of main focuses in this work is to develop ANN models for daily stream flow forecasting and determine a suitable combination of input variables and a more accurate architecture in the design phase. Another focus is to compare the performance of ANN models and TOPMODEL in one day ahead stream flow forecasting. Baohe River basin, with a humid climate, is selected as the study area. The results show that ANN models with flow data plus precipitation data as the input variables perform much better than that with only precipitation data or only flow data as the input variables. The performance of ANN models will be slightly reduced if evaporation data are added into the input vector. ANN has a very good performance against the TOPMODEL in terms of Nash-Sutcliffe efficiency. Nevertheless, they both can not capture the main peak flow: ANN underestimates the main peak flows while TOPMODEL overestimates two or three peak flows in validation years.
Improving forecasting accuracy of medium and long-term runoff using artificial neural network based on EEMD decomposition

Abstract:Hydrological time series forecasting is one of the most important applications in modern hydrology, especially for the effective reservoir management. In this research, an artificial neural network (ANN) model coupled with the ensemble empirical mode decomposition (EEMD) is presented for forecasting medium and long-term runoff time series. First, the original runoff time series is decomposed into a finite and often small number of intrinsic mode functions (IMFs) and a residual series using EEMD technique for attaining deeper insight into the data characteristics. Then all IMF components and residue are predicted, respectively, through appropriate ANN models. Finally, the forecasted results of the modeled IMFs and residual series are summed to formulate an ensemble forecast for the original annual runoff series. Two annual reservoir runoff time series from Biuliuhe and Mopanshan in China, are investigated using the developed model based on four performance evaluation measures (RMSE, MAPE, R and NSEC). The results obtained in this work indicate that EEMD can effectively enhance forecasting accuracy and the proposed EEMD-ANN model can attain significant improvement over ANN approach in medium and long-term runoff time series forecasting.
Daily Streamflow Forecasting by Artificial Neural Network in a Large-Scale Basin

Abstract:Artificial Neural Network (ANN) models have been successfully applied to daily stream flow forecasting in many basins. However, most of them are designed for small or meso-scale basins rather than large-scale basins. One of aims in this work is to develop an ANN model with an optimized combination of input variables and a more accurate architecture for daily stream flow forecasting. Another aim is to compare the performance of ANN models and a rainfall-runoff model—XXT, which is a new efficient hybrid model of Xinanjiang model and TOPMODEL, in one day in advance stream flow forecasting. Yingluoxia basin, with a drainage area of 10009 km2, is chosen as a large-scale basin. The results show that the stream flow, precipitation and evaporation are all necessary to ANN modeling for this basin. The ANN model with an appropriate combination of stream flow, precipitation and evaporation as input vector performs much better than XXT in terms of Nash-Sutcliffe efficiency. Even if only using antecedent stream flow data as inputs ANN models are still better than XXT model for one day in advance flow forecasting.
Runoff Prediction of Bharathapuzha River Basin using Artificial Neural Network and SWAT Model

Abstract:An attempt was made to model the non-linear system of rainfall-runoff process from Bharathapuzha River basin using an information processing paradigm, Artificial Neural Network (ANN). The results were compared with the outputs of the semi-distributed, physically-based SWAT (Soil and Water Assessment Tool) model. The ANN modelling was done using back propagation learning algorithm, tan sigmoid transfer function, and model input strategy having rainfall and other climatic variables as input by assigning number of layers as 5, 10, 15, 20, 25, 30, and 40. Different models were evaluated with respect to coefficient of correlation (r), coefficient of determination (R2 ), and root mean square error (RMSE). Among the ANN models, ANN-BP-A-5 (six input variables, 5 hidden layers) performed best, followed by ANN-BP-A40 (six input variables, 40 hidden layers). Comparison of ANN predicted runoff of the best models (ANN-BP-A-5 and ANNBP-A40) with the SWAT predicted runoff revealed that the simulated runoff using SWAT was more correlated to observed runoff than ANN predicted runoff. The ANN models underestimated the flow during the rainy season, and gave an overestimation during the summer season. However, the R2 values of 0.666 and 0.649 obtained for ANN-BP-A-5 and ANN-BP-A40, respectively, indicated that the performances of ANN models were satisfactory and ANN model can also be used for runoff prediction in data scarce areas.

Abstract:The important foundation for water resource management and utilization is effective monthly runoff prediction. In this study, a new coupled model for predicting monthly runoff is proposed. In order to predict the decomposed subsequences separately using an ELMAN neural network optimized by the sparrow search algorithm (SSA), this model first decomposes the original runoff series using robust local mean decomposition (RLMD) and complete ensemble empirical mode decomposition with adaptive noise (CEEMDAN) predicts the decomposed subsequences separately using an ELMAN neural network optimized by the sparrow search algorithm (SSA), and reconstructs the results to get initial prediction results. To acquire the final prediction result, local error correction (LEC) is used to perform error correction on the initial prediction model. Five evaluation indicators are used to assess the performance of the suggested coupling model on monthly runoff data from three experimental stations in China. After having analyzed the error correction capability of LEC model, it is found that CEEMDAN-RLMD-SSA-ELMAN-LEC decreases root mean square error (RMSE) values of Manwan Hydropower, Jiayuguan Station, and Yingluoxia Station by 18.52%, 21.78%, and 38.80%, respectively, and increases Nash-Sutcliffe efficiency coefficient (NSEC) values by 2.11%, 4.49%, and 5.43% compared to CEEMDAN-RLMD-SSA-ELMAN without error correction. Therefore, by incorporating error correction, the proposed coupled model is a trustworthy and beneficial means for forecasting monthly runoff.

Abstract:A forecasting model is developed using a hybrid approach of artificial neural network (ANN) and multiple regression analysis (MRA) to predict the total typhoon rainfall and groundwater-level change in the Zhuoshui River basin. We used information from the raingauge stations in eastern Taiwan and open source typhoon data to build the ANN model for forecasting the total rainfall and the groundwater level during a typhoon event; then we revised the predictive values using MRA. As a result, the average accuracy improved up to 80% when the hybrid model of ANN and MRA was applied, even where insufficient data were available for model training. The outcome of this research can be applied to forecasts of total rainfall and groundwater-level change before a typhoon event reaches the Zhuoshui River basin once the typhoon has made landfall on the east coast of Taiwan.
