Abstract:FY-2C is a geo-stationary orbiting meteorological satellite designed by China independently. Based on statistical and spectral analysis of FY-2C data, this paper proposed a new cloud detection index operating accurately and quickly in spite of the low spatial resolution few spectral information. The diversity and sensitivity of cloud for each of the 4 bands of FY-2C data is also analyzed in this paper. The Infrared Red band 1, band 3 is found to be most suitable for cloud detection due to their spectral sensitivity of cloud.

Abstract:Cloud cover is an important issue for Earth observation satellite imaging. When the proportion of clouds in the remote sensing image is too high,or the specific target is not visible,the remote sensing image will be invalid. Earth observation satellites can choose among multiple observation targets based on cloud forecast information. For the application of Earth observation satellite mission planning, a large-area short-term cloud forecasting method was proposed. First, the cloud motion vector was obtained by the Farneback optical flow method. Subsequently, the predicted cloud image can be obtained by extrapolating the cloud motion vector. Meanwhile, the Laplace operator was introduced to depict the characterization of the diffusion phenomenon in the process of cloud movement. Utilizing the real cloud image sequence data of the FY -2 satellite, the diffusion factor can be optimized through the backpropagation algorithm of the neural network to improve the effect of cloud forecasting. Through the analysis of forecasting results, the introduced Laplace operator method can improve the accuracy of cloud forecasting. The error of the 80% quantile of cloud coverage is about 11.7%. The cloud cover forecasting with this level of accuracy can be used to guide the mission planning of Earth observation satellites.

Abstract:The spectral area ratio method (SARM ) was proposed to detect clouds from Landsat 8 images . Landsat 8 visible to near infrared bands (band 1-band 5) and thermal infrared bands (band 10-band 11) were used based on spectral analysis on clouds and other ground objects in order to establish pixels-based spectral area ratio .Scatter plot for images was plotted with normalized difference vegetation index (NDVI) and spectral area ratio .Clouds were detected with different confidence intervals (high ,medium and low level).Three Landsat 8 images of different spatial were employed to demonstrate the accuracy of the method with three representative zones from each image and 10 000 pixels from each zone.Results show that spectral area ratio can enhance the difference between clouds and underlying surface , which is beneficial for the cloud detection .Scatter plot based on NDVI and spectral area ratio can clearly display the cloud distribution features under different ground conditions . The extraction method of adjustable threshold can meet requirements of cloud detection with various objectives .The method can significantly improve the overall accuracy by 10% compared with three previous cloud detection methods .

Abstract:A variety of clouds are present in almost all moderate-resolution imaging spectroradiometer (MODIS) images. To extract accurate information from MODIS data, a key preprocessing step is to detect the cloudy pixels. This article proposes a new algorithm to distinguish between cloudy and cloud-free pixels in MODIS images. This algorithm is based on the differences in the spectral areas between clouds and other surface features. It uses as many as 24 of the 36 MODIS spectral bands to obtain the integrated spectral information. The method has been illustrated by an example of 76 MODIS images recorded from 2011 to 2013. The results show that the algorithm is capable of correctly identifying most of the cloud-contaminated pixels except for some thin cloud pixels. We compared the new method with the MODIS Cloud Mask algorithm and found that the new algorithm performs better than the MODIS MOD35 Cloud Mask in some situation, such as coastal area, sun glint, and data with invalid values. Pour extraire des informations precises a partir des donnees MODIS, une etape cle de pretraitement est de detecter les pixels nuageux. Cet article propose un nouvel algorithme pour distinguer les pixels avec nuages des pixels sans nuages dans les images MODIS. Cet algorithme est base sur les differences dans les zones du spectre entre les nuages et d'autres caracteristiques de surface. Il utilise jusqu'a 24 des 36 bandes spectrales de MODIS pour obtenir les informations spectrales integrees. La methode a ete illustree sur un echantillon de 76 images MODIS prises entre 2011 et 2013. Les resultats montrent que l'algorithme est capable d'identifier correctement la plupart des pixels contamines par les nuages a l'exception de quelques pixels avec des nuages minces. Nous avons compare la nouvelle methode avec l'algorithme pour le masquage des nuages de MODIS et nous avons constate que le nouvel algorithme est plus performant que le masque des nuages MOD35 de MODIS dans certaines situations, comme dans les zones cotieres, pour la zone du reflet solaire et pour les donnees avec des valeurs non valides.

Abstract:Cloud obscuration in remote sensing images affects Earth observation tasks by causing blurred and incomplete surface observation information. Regarding this, cloud detection is crucial in the processing of remote sensing images. However, existing cloud detection methods present some challenges, such as missed detection of thin cloud areas and false detection caused by confusing clouds with highlighted areas such as snow and ice. To address these problems, in this article, we proposed a cloud detection network that incorporates spectral feature enhancement and spatial-spectral feature fusion. Based on the difference in reflectivity of clouds and ground objects in the atmosphere, we proposed a short-wave infrared cloud index (SWIR-Index) and designed a feature-guided module to incorporate the spectral feature into the network and guide the training of the network to enhance the network's ability to learn differential features of snow, ice, and clouds. To fully utilize the spectral band information and spatial features of remote sensing images, we developed a spatial-spectral feature fusion module (SSFFM) that extracts spatial features at different scales and performs inter-spectral information fusion of spectral bands. Furthermore, we proposed a encoder-decoder feature fusion module that automatically calculates pixel weights by using a weight extraction block. The ablation study proves that our method can improve the feature extraction ability, reduce the leakage and misdetection, and improve the detection accuracy. Experimental results on Sentinel-2A images demonstrate the superior performance of the method, reaching 98.65(%) overall accuracy (OA) on the WHUS2-CD dataset, 97.50(%) on the S2-CMC dataset, and 92.36(%) on the CloudSEN12 dataset, which outperforms other algorithms.

Abstract:The rapid cloud detection method in various backgrounds is studied based on the spectral reflection characteristics. The spectral reflection characteristics are combined with the texture features of the clouds, and a comprehensive cloud detection algorithm is proposed based on the combination of dynamic fractal dimension and radiation quantity characteristics. The hyperspectral remote sensing images taken by the Hyperion sensor of the EO-1 satellite are taken as examples to study the cloud-containing remote sensing images of different underlying surfaces, and the thick clouds area and thin clouds area are detected and analyzed. Compared with the two algorithms of remote sensing image cloud detection, the proposed algorithm can identify the thin cloud regions more accurately, which can greatly improve the accuracy of remote sensing image cloud detection and at the same time can meet the requirements of fast cloud detection of satellite-borne hyperspectral images.

Abstract:Basic clustering algorithms including K-means, fusion c-means and C4.5 decision tree have been applied in cloud detection with FY-2C data. With the limitation that no reliable template is available, supervised classification algorithm is utilized to test the credibility of non-supervised classification algorithms, which contribute to generate a cloud classification model with high credibility. It is proved that cloud classification product distributed by National Satellite Meteorological Center enjoys a high credibility and stability. It is also demonstrated that FY-2C data is eligible to classify cloud into 4 types as cumulonimbus, cirrostratus, dense-cirrus and low and middle cloud.

Abstract:Clouds are a very important factor in the availability of optical remote sensing images. Recently, deep learning (DL)-based cloud detection methods have surpassed classical methods based on rules and physical models of clouds. However, most of these deep models are very large, which limits their applicability and explainability, while other models do not make use of the full spectral information in multispectral images, such as Sentinel-2. In this article, we propose a lightweight network for cloud detection, fusing multiscale spectral and spatial features (CD-FM3SFs) and tailored for processing all spectral bands in Sentinel-2A images. The proposed method consists of an encoder and a decoder. In the encoder, three input branches are designed to handle spectral bands at their native resolution and extract multiscale spectral features. Three novel components are designed: a mixed depthwise separable convolution (MDSC) and a shared and dilated residual block (SDRB) to extract multiscale spatial features, and a concatenation and sum (CS) operation to fuse multiscale spectral and spatial features with little calculation and no additional parameters. The decoder of CD-FM3SF outputs three cloud masks at the same resolution as input bands to enhance the supervision information of small, middle, and large clouds. To validate the performance of the proposed method, we manually labeled 36 Sentinel-2A scenes evenly distributed over mainland China. The experiment results demonstrate that CD-FM3SF outperforms traditional cloud detection methods and state-of-the-art DL-based methods in both accuracy and speed.

Abstract:Cloud detection is a fundamental step for optical satellite image applications. Existing deep learning methods can provide more accurate cloud detection results. However, the performance of these methods relies on a large number of label samples, whose collection is time-consuming and high-cost. In addition, cloud detection is challenging in high-brightness scenes due to cloud and high-brightness objects having a similar spectral features. In this study, we propose a cloud index driven spectral-spatial-context attention network (SSCA-net) for cloud detection, which relies on no effort to manually collect label samples and can improve the accuracy of cloud detection in high-brightness scenes. The label samples are automatically generated from the cloud index by using dual-threshold, which is then expanded to improve the completeness of cloud mask labels. We designed SSCA-net with the spectral-spatial-context aware module and spectral-spatial-context information aggregation module, aimed to improve the accuracy of cloud detection in high-brightness scenes. The results show that the proposed SSCA-net achieved good performance with an average overall accuracy of 97.69% and an average kappa coefficient of 92.71% on the Sentinel-2 and Landsat-8 datasets. This article provides fresh insight into how advanced deep attention networks and cloud indexes can be integrated to obtain high accuracy of cloud detection on high-brightness scenes.

Abstract:Double-layer cloud is a special cloud condition, and clouds in two layers have different effects on solar radiation reaching ground. Getting the shape of double-layer clouds is helpful to study the change of solar irradiance. The proposed double-layer clouds detection method is based on the cloud base height (CBH) and brightness of double-layer clouds. The CBH is calculated based on binocular parallax, which requires two images filmed synchronously by two cameras, and the brightness is offered by the brightness channel in HSV color space. The accuracy of this method is 98.5% for single-layer clouds and 89.4% for double-layer clouds. The reasons for misidentifications are (1) the brightness contrast decreases when the high-layer clouds are thick, (2) the distant low clouds have different brightness in top and bottom.

Abstract:There are challenges for cloud detection over bright surfaces, especially for Sentinel-2 image without thermal band. In this paper, we developed a new cloud detection algorithm for Sentinel-2 data designed to tackle the challenges of cloud detection on bright targets. Our algorithm (called RF-NDTeI-SNIC) was built through the integration of Random Forest (RF) model, Normalized Difference Temporal Index (NDTeI) cloud index and Simple Non-Iterative Clustering (SNIC) image segmentation algorithm. First, RF and NDTeI were used to derive the initial and second stage's cloud detection results, respectively. Then, the RF- and NDTeI-based results were fused to remove the bright surfaces and land cover changes. Finally, the fusion results were further refined using SNIC for morphological processing. The proposed RF-NDTeI-SNIC algorithm was evaluated using nine challenging cloud-covered Sentinel-2 scenes with substantial bright surfaces. Results indicated that the average overall accuracy of our algorithm was 95.01%, with average commission rate of 10.19% for cloud. In addition, five commonly used Sentinel-2 cloud mask algorithms including s2cloudless, QA, Fmask, CDI and Tmask were selected for comparative analysis. Results suggested that our algorithm outperformed others with overall accuracies of 89.60–94.17% and cloud commission rate of 9.46–37.50%, and have significant advantages in terms of bright surfaces. In summary, the RF-NDTeI-SNIC algorithm we developed was capable of yielding accurate Sentinel-2 cloud masks, and the novel NDTeI cloud index we proposed gave a new and effective approach for improving the separability of clouds and bright surfaces.

A Cloud Detection Algorithm Based on FY-4A/GIIRS Infrared Hyperspectral Observations

Abstract:Cloud detection is an essential preprocessing step when using satellite-borne infrared hyperspectral sounders for data assimilation and atmospheric retrieval. In this study, we propose a cloud detection algorithm based solely on the sensitivity and detection characteristics of the FY-4A Geostationary Interferometric Infrared Sounder (GIIRS), rather than relying on other instruments. The algorithm consists of four steps: (1) combining observed radiation and clear radiance data simulated by the Community Radiative Transfer Model (CRTM) to identify clear fields of view (FOVs); (2) determining the number of clouds within adjacent 2 × 2 FOVs via a principal component analysis of observed radiation; (3) identifying whether there are large observed radiance differences between adjacent 2 × 2 FOVs to determine the mixture of clear skies and clouds; and (4) assigning adjacent 2 × 2 FOVs as a cloud cluster following the three steps above to select an appropriate classification threshold. The classification results within each cloud detection cluster were divided into the following categories: clear, partly cloudy, or overcast. The proposed cloud detection algorithm was tested using one month of GIIRS observations from May 2022 in this study. The cloud detection and classification results were compared with the FY-4A Advanced Geostationary Radiation Imager (AGRI)'s operational cloud mask products to evaluate their performance. The results showed that the algorithm's performance is significantly influenced by the surface type. Among all-day observations, the highest recognition performance was achieved over the ocean, followed by land surfaces, with the lowest performance observed over deep inland water. The proposed algorithm demonstrated better clear sky recognition during the nighttime for ocean and land surfaces, while its performance was higher for partly cloudy and overcast conditions during the day. However, for inland water surfaces, the algorithm consistently exhibited a lower cloud recognition performance during both the day and night. Moreover, in contrast to the GIIRS's Level 2 cloud mask (CLM) product, the proposed algorithm was able to identify partly cloudy conditions. The algorithm's classification results departed slightly from those of the AGRI's cloud mask product in areas with clear sky/cloud boundaries and minimal convective cloud coverage; this was attributed to the misclassification of clear sky as partly cloudy under a low-resolution situation. AGRI's CLM products, temporally and spatially collocated to the GIIRS FOV, served as the reference value. The proportion of FOVs consistently classified as partly cloudy to the total number of partly cloudy FOVs was 40.6%. In comparison with the GIIRS's L2 product, the proposed algorithm improved the identification performance by around 10%.

Abstract:For optical remote sensing images with high spatial resolution and low spectral number, the complexity of ground objects poses great challenges to cloud detection algorithms, such as the differentiation of clouds from objects with similar features as clouds and the identification of thin clouds. In this paper, a novel cloud detection method is proposed for Gaofen-2 remote sensing imagery. The radiation transmittance is estimated based on the dark channel prior, and the overestimated radiation transmittance is corrected using spectral features. A three-step post-processing strategy is adopted to eliminate misidentification introduced by the highlighted surfaces based on object geometric, textural, and boundary features. In the experiments, Gaofen-2 multispectral images with different cloud categories and cloud thicknesses are involved to evaluate the performance of the proposed method. The results show that the proposed method can obtain an average cloud detection accuracy of 0.9573 on six different clouds. The proposed algorithm can also effectively detect both thick and thin clouds with an average accuracy of more than 0.9517. The advantages of the method for thin cloud detection are further demonstrated by comparison with existing algorithms.

Abstract:Cloud macro and micro physical characteristic parameters play an important role not on-ly in the field of the analysis and forecast of the weather and climate, but also in the field of weather modification to identify the seeding condition. Based on the data from FY-2C/D stationary satellite and SBDART radiation transfer model, associated with the sounding data and surface information, a method retrieving cloud macro and micro physical parameters is established in this research. These parameters include cloud top height, cloud top temperature, depth of super-cooled layer, depth of warm layer, cloud bottom height, depth of cloud, cloud optical thickness, cloud effective particle radius and cloud liquid water content. It has been run operationally. In this paper, the correlated information such as physical meaning, retrieving method and technology, retrieving process and data format are simply introduced. Furthermore, comparing with the observation of Cloudsat up to the minute, the retrieving results of main cloud parameters are proved to be reasonable and usable. By contrast with same kind products of MODIS, it also shows good corresponding relationship.
Operational application of Fengyun geostationary meteorological satellites to cloud observation products

Abstract:Cloud products from geostationary satellites are the main alternative to surface synoptic cloud observations (SYNOP), and have become the baseline products for the development and construction of the Quality Management System (QMS) of integrated meteorological observation in China. This study addresses the needs of the China Meteorological Administration (CMA) for such an operational reform, and it is carried out using real-time observations obtained from the Fengyun-2E (FY-2E) geostationary satellite in 2012 to derive cloud total amount and classification using two different methods. Compared to surface SYNOP observations, the cloud total amount estimated by FY-2E is generally significantly lower (about 30% lower on average). The cloud classification resulting from the two methods used in this study is also significantly different from the classification obtained from surface observations (difference between 22 and 32%). The difference is smaller for the classification method, which uses additional auxiliary temperature profiles.
A Cloud Detection Method for Vertically Pointing Millimeter-Wavelength Cloud Radar

Abstract:A new method using three dimensions of cloud continuity, including range dimension, Doppler dimension, and time dimension, is proposed to discriminate cloud from noise and detect more weak cloud signals in vertically pointing millimeter-wave cloud radar observations by fully utilizing the spatiotemporal continuum of clouds. A modified noise level estimation method based on the Hildebrand and Sekhon algorithm is used for more accurate noise level estimation, which is critical for weak signals. The detection method consists of three steps. The first two steps are performed at the Doppler power spectrum stage, while the third step is performed at the base data stage. In the first step, a new adaptive spatial filter combined with the Kuwaraha filter and the Gaussian filter, using the ratio of mean to standard deviation as the adaptive parameter, is applied to initially mask the potential cloud signals to improve the detection performance at the boundary of cloud and noise. Simulations of boundary cases were performed to compare our adaptive filter and normal Gaussian filters. Box filters are used in steps two and three to remove the remaining noise. We applied our method to cloud radar observations with TJ-II cloud radar at the Nanjing University of Information Science & Technology. The results showed that our method can detect more weak cloud signals than the usual methods, which are performed only at the Doppler power spectrum stage or the base data stage.

Abstract:A method of hydrometeor detection using CLOUDSAT data is described.To solve the problem of fuzzy cloud edge and to maintain most edge information,a way of edge detection using wavelet transform is presented to detect cloud edge.The method acquires the information of the cloud edge by detecting the image local maxima of the two-dimension wavelet transform.The algorithm was verified by a brief comparison between experiment results and the results achieved by CLOUDSAT project using SEM(Significant Echo Mask)algorithm.

Abstract:Nowadays, GF-1 (GF is the acronym for GaoFen which means high-resolution in Chinese) remote sensing images are widely utilized in agriculture because of their high spatio-temporal resolution and free availability. However, due to the transferrable rationale of optical satellites, the GF-1 remote sensing images are inevitably impacted by clouds, which leads to a lack of ground object's information of crop areas and adds noises to research datasets. Therefore, it is crucial to efficiently detect the cloud pixel of GF-1 imagery of crop areas with powerful performance both in time consumption and accuracy when it comes to large-scale agricultural processing and application. To solve the above problems, this paper proposed a cloud detection approach based on hybrid multispectral features (HMF) with dynamic thresholds. This approach combined three spectral features, namely the Normalized Difference Vegetation Index (NDVI), WHITENESS and the Haze-Optimized Transformation (HOT), to detect the cloud pixels, which can take advantage of the hybrid Multispectral Features. Meanwhile, in order to meet the variety of the threshold values in different seasons, a dynamic threshold adjustment method was adopted, which builds a relationship between the features and a solar altitude angle to acquire a group of specific thresholds for an image. With the test of GF-1 remote sensing datasets and comparative trials with Random Forest (RF), the results show that the method proposed in this paper not only has high accuracy, but also has advantages in terms of time consumption. The average accuracy of cloud detection can reach 90.8% and time consumption for each GF-1 imagery can reach to 5 min, which has been reduced by 83.27% compared with RF method. Therefore, the approach presented in this work could serve as a reference for those who are interested in the cloud detection of remote sensing images.
A Novel Classification Extension-Based Cloud Detection Method for Medium-Resolution Optical Images

Abstract:Accurate cloud detection using medium-resolution multispectral satellite imagery (such as Landsat and Sentinel data) is always difficult due to the complex land surfaces, diverse cloud types, and limited number of available spectral bands, especially in the case of images without thermal bands. In this paper, a novel classification extension-based cloud detection (CECD) method was proposed for masking clouds in the medium-resolution images. The new method does not rely on thermal bands and can be used for masking clouds in different types of medium-resolution satellite imagery. First, with the support of low-resolution satellite imagery with short revisit periods, cloud and non-cloud pixels were identified in the resampled low-resolution version of the medium-resolution cloudy image. Then, based on the identified cloud and non-cloud pixels and the resampled cloudy image, training samples were automatically collected to develop a random forest (RF) classifier. Finally, the developed RF classifier was extended to the corresponding medium-resolution cloudy image to generate an accurate cloud mask. The CECD method was applied to Landsat-8 and Sentinel-2 imagery to test the performance for different satellite images, and the well-known function of mask (FMASK) method was employed for comparison with our method. The results indicate that CECD is more accurate at detecting clouds in Landsat-8 and Sentinel-2 imagery, giving an average F-measure value of 97.65% and 97.11% for Landsat-8 and Sentinel-2 imagery, respectively, as against corresponding results of 90.80% and 88.47% for FMASK. It is concluded, therefore, that the proposed CECD algorithm is an effective cloud-classification algorithm that can be applied to the medium-resolution optical satellite imagery.

Abstract:Multilayer cloud system, such as density cirrus, thin cirrus cloud overlaying a low-level water cloud and density water cloud was detected by using bispectral methods that scatter plot of the near-infrared 1.6 mum channel reflectance and the 11 mum brightness temperatures and brightness temperature difference between 3.75 mum and 11 mum channel data from FY-1D and NOAA. Results show that the methods have a promising facility for identifying areas containing typical multilayer cloud system by multi channel data.
