Thus mining networks by assuming only one kind of relation may miss a lot of valuable hidden community information and may not be adaptable to the diverse information needs from different users.In this paper, we systematically analyze the problem of mining hidden communities on heterogeneous social networks. Based on the observation that different relations have different importance with respect to a certain query, we propose a new method for learning an optimal linear combination of these relations which can best meet the user's expectation. With the obtained relation, better performance can be achieved for community mining. Our approach to social network analysis and community mining represents a major shift in methodology from the traditional one, a shift from single-network, user-independent analysis to multi-network, user-dependant, and query-based analysis. Experimental results on Iris data set and DBLP data set demonstrate the effectiveness of our method.

Abstract:In reality, there exist multiple heterogeneous social networks, each representing a particular kind of relationship, and each kind of relationship may play a distinct role in a particular task. It is unsuitable to assume only one kind of relation in mining community. Recently, a new relation extraction algorithm was proposed. However, this method fails to handle the indirect relation which exists generally. This paper investigates this problem and proposes several methods to mine heterogeneous social networks with indirect connecting. The experiments on the DBLP data sets validate the effectiveness of our method.

Abstract:Community is a common characteristic of networks including social networks, biological networks, computer and information networks, to name a few. Community detection is a basic step for exploring and analysing these network data. Typically, homogenous network is a type of networks which consists of only one type of objects with one type of links connecting them. There has been a large body of developments in models and algorithms to detect communities over it. However, real-world networks naturally exhibit heterogeneous qualities appearing as multiple types of objects with multi-relational links connecting them. Those heterogeneous information could facilitate the community detection for its constituent homogeneous networks, but has not been fully explored. In this paper, we exploit heterogeneous multi-relational networks (HMRNet) and propose an efficient message passing based algorithm to simultaneously detect communities for all homogeneous networks. Specifically, an HMRNet is reorganized into a hierarchical structure with homogeneous networks as its layers and heterogeneous links connecting them. To detect communities in such an HMRNet, the problem is formulated as a maximum a posterior (MAP) over a factor graph. Finally a message passing based algorithm is derived to find a best solution of the MAP problem. Evaluation on both synthetic and real-world networks confirms the effectiveness of the proposed method.

Abstract:Heterogeneous graph representation techniques can be applied in many real-world applications. Even the natural languages that are usually modeled as sequential data can also be constructed as a heterogeneous graph by some techniques, so as to widely and accurately capture the complex interactions among the words, entities, topics, instances, and other components of the texts. In this chapter, we focus on summarizing the heterogeneous graph representation applications on text mining. Particularly, we introduce several heterogeneous graph based text mining methods, including HGAT for short text classification, GUND and GNewsRec for news recommendation. In the field of heterogeneous graph representation for text mining, methods mainly contain two key components: heterogeneous graph construction from texts and heterogeneous graph representation algorithm for tasks. We will roughly illustrate heterogeneous graph modeling for text mining tasks from these two points.

Abstract:In social networks, users and artifacts (documents, discussions or videos) can be modelled as directed bi-type heterogeneous networks. Most existing works for community detection is either with undirected links or in homogeneous networks. In this paper, we propose an efficient algorithm OcdRank (Overlapping Community Detection and Ranking), which combines overlapping community detection and community-member ranking together in directed heterogeneous social network. The algorithm has low time complexity and supports incremental update. Experiments show that our method can detect better community structures as compared to other existing community detection methods.

Abstract:Social media networks are playing increasingly prominent role in people’s daily life. Community structure is one of the salient features of social media network and has been applied to practical applications, such as recommendation system and network marketing. With the rapid expansion of social media size and surge of tremendous amount of information, how to identify the communities in big data scenarios has become a challenge. Based on our previous work and the map equation (an equation from information theory for community mining), we develop a novel distributed community structure mining framework. In the framework, (1) we propose a new link information update method to try to avoid data writing related operations and try to speedup the process. (2) We use the local information from the nodes and their neighbors, instead of the pagerank, to calculate the probability distribution of the nodes. (3) We exclude the network partitioning process from our previous work and try to run the map equation directly on MapReduce. Empirical results on real-world social media networks and artificial networks show that the new framework outperforms our previous work and some well-known algorithms, such as Radetal, FastGN, in accuracy, velocity and scalability.

Abstract:Mining different types of communities from web data have attracted a lot of research efforts in recent years. However, none of the existing community mining techniques has taken into account both the dynamic as well as heterogeneous nature of web data. In this paper, we propose to characterize and predict community members from the evolution of heterogeneous web data. We first propose a general framework for analyzing the evolution of heterogeneous networks. Then, the academic network, which is extracted from 1 million computer science papers, is used as an example to illustrate the framework. Finally, two example applications of the academic network are presented. Experimental results with a real and very large heterogeneous academic network show that our proposed framework can produce good results in terms of community member recommendation. Also, novel knowledge and insights can be gained by analyzing the community evolution pattern.

Abstract:Detecting and monitoring competitors is fundamental to a company to stay ahead in the global market. Existing studies mainly focus on mining competitive relationships within a single data source, while competing information is usually distributed in multiple networks. How to discover the underlying patterns and utilize the heterogeneous knowledge to avoid biased aspects in this issue is a challenging problem. In this paper, we study the problem of mining competitive relationships by learning across heterogeneous networks. We use Twitter and patent records as our data sources and statistically study the patterns behind the competitive relationships. We find that the two networks exhibit different but complementary patterns of competitions. Our proposed model, Topical Factor Graph Model (TFGM), defines a latent topic layer to bridge the two networks and learns a semi-supervised learning model to classify the relationships between entities (e.g., companies or products). We test the proposed model on two real data sets and the experimental results validate the effectiveness of our model, with an average of +46\% improvement over alternative methods.

Abstract:The community plays a crucial role in understanding user behavior and network characteristics in social networks. Some users can use multiple social networks at once for a variety of objectives. These users are called overlapping users who bridge different social networks. Detecting communities across multiple social networks is vital for interaction mining, information diffusion, and behavior migration analysis among networks. This paper presents a community detection method based on nonnegative matrix tri-factorization for multiple heterogeneous social networks, which formulates a common consensus matrix to represent the global fused community. Specifically, the proposed method involves creating adjacency matrices based on network structure and content similarity, followed by alignment matrices which distinguish overlapping users in different social networks. With the generated alignment matrices, the method could enhance the fusion degree of the global community by detecting overlapping user communities across networks. The effectiveness of the proposed method is evaluated with new metrics on Twitter, Instagram, and Tumblr datasets. The results of the experiments demonstrate its superior performance in terms of community quality and community fusion.

Significant-attributed Community Search in Heterogeneous Information Networks

Abstract:Community search is a personalized community discovery problem aimed at finding densely-connected subgraphs containing the query vertex. In particular, the search for communities with high-importance vertices has recently received a great deal of attention. However, existing works mainly focus on conventional homogeneous networks where vertices are of the same type, but are not applicable to heterogeneous information networks (HINs) composed of multi-typed vertices and different semantic relations, such as bibliographic networks. In this paper, we study the problem of high-importance community search in HINs. A novel community model is introduced, named heterogeneous significant community (HSC), to unravel the closely connected vertices of the same type with high attribute values through multiple semantic relationships. An HSC not only maximizes the exploration of indirect relationships across entities of the anchor-type but incorporates their significance. To search the HSCs, we first develop online algorithms by exploiting both segmented-based meta-path expansion and significance increment. Specially, a solution space reuse strategy based on structural nesting is designed to boost the efficiency. In addition, we further devise a two-level index to support searching HSCs in optimal time, based on which a space-efficient compact index is proposed. Extensive experiments on real-world large-scale HINs demonstrate that our solutions are effective and efficient for searching HSCs, and the index-based algorithms are 2-4 orders of magnitude faster than online algorithms.

Abstract:ABSTRACTInfluence is a complex and subtle force that governs the dynamics of social networks as well as the behaviors of involved users. Understanding influence can benefit various applications such as viral marketing, recommendation, and information retrieval. However, most existing works on social influence analysis have focused on verifying the existence of social influence. Few works systematically investigate how to mine the strength of direct and indirect influence between nodes in heterogeneous networks. To address the problem, we propose a generative graphical model which utilizes the heterogeneous link information and the textual content associated with each node in the network to mine topic-level direct influence. Based on the learned direct influence, a topic-level influence propagation and aggregation algorithm is proposed to derive the indirect influence between nodes. We further study how the discovered topic-level influence can help the prediction of user behaviors. We validate the approach on three different genres of data sets: Twitter, Digg, and citation networks. Qualitatively, our approach can discover interesting influence patterns in heterogeneous networks. Quantitatively, the learned topic-level influence can greatly improve the accuracy of user behavior prediction.
Learning a Probabilistic Semantic Model from Heterogeneous Social Networks for Relationship Identification

Abstract:Nowadays, social networks play an important role in our lives, in which information and knowledge are exchanged, shared and transformed. With time, large volumes of real-world data have been accumulated capturing diversified application domains. However, heterogeneity and incompleteness of data make social networks perform as 'data isolated islands' separated to each other. In this paper, we propose a generic approach that consists of an ontology-based social network integration approach and a statistic learning method towards the Semantic Web data. In particular, an extended FOAF (Friend-Of-A-Friend) ontology is used as the mediation schema to integrate social networks and a hybrid entity reconciliation method is used to resolve entities of different data sources. We also present an analyzing approach that learns a probabilistic semantic model (PSM) from social data for relationship identification. Empirical results prove that, compared with single numeric or logical methods respectively, our hybrid reconciliation method has obvious improvements on precision and recall during combining LinkedIn.com and DBLP. In addition, PSM framework can reserve richer semantics of semantic data completely during data analysis.

Abstract:Citation relationship between scientific publications has been successfully used for scholarly bibliometrics, information retrieval and data mining tasks, and citation-based recommendation algorithms are well documented. While previous studies investigated citation relations from various viewpoints, most of them share the same assumption that, if paper 1 cites paper 2 (or author 1 cites author 2 ), they are connected, regardless of citation importance, sentiment, reason, topic, or motivation. However, this assumption is oversimplified. In this study, we employ an innovative “context-rich heterogeneous network” approach, which paves a new way for citation recommendation task. In the network, we characterize (1) the importance of citation relationships between citing and cited papers, and (2) the topical citation motivation. Unlike earlier studies, the citation information, in this paper, is characterized by citation textual contexts extracted from the full-text citing paper. We also propose algorithm to cope with the situation when large portion of full-text missing information exists in the bibliographic repository. Evaluation results show that, context-rich heterogeneous network can significantly enhance the citation recommendation performance.
A Concentric-Circle Model for Community Mining in Graph Structures

Abstract:Discovering communities from a graph structure such as the Web has become an interesting research problem recently. In this paper, comparing with the state-of-the-art authority detecting and graph partitioning methods, we propose a concentric-circle model to more accurately define communities. With this model, a community could be described as a set of concentric-circles. The most important objects representing the concept of a whole community lie in the center and are called core objects. Affiliated objects, which are related to the core objects, surround the core with different ranks. Base on the concentric-circle model, a novel algorithm is developed to discover communities conforming to this model. We also conducted a case study to automatically discover research interest groups in the computer science domain from the Web. Experiments show that our method is very effective to generate high-quality communities with more clear structure and more tunable granularity.

Abstract:Every piece of textual data is generated as a method to convey its authors' opinion regarding specific topics. Authors deliberately organize their writings and create links, i.e., references, acknowledgments, for better expression. Thereafter, it is of interest to study texts as well as their relations to understand the underlying topics and communities. Although many efforts exist in the literature in data clustering and topic mining, they are not applicable to community discovery on large document corpus for several reasons. First, few of them consider both textual attributes as well as relations. Second, scalability remains a significant issue for large-scale datasets. Additionally, most algorithms rely on a set of initial parameters that are hard to be captured and tuned. Motivated by the aforementioned observations, a hierarchical community model is proposed in the paper which distinguishes community cores from affiliated members. We present our efforts to develop a scalable community discovery solution for large-scale document corpus. Our proposal tries to quickly identify potential cores as seeds of communities through relation analysis. To eliminate the influence of initial parameters, an innovative attribute-based core merge process is introduced so that the algorithm promises to return consistent communities regardless initial parameters. Experimental results suggest that the proposed method has high scalability to corpus size and feature dimensionality, with more than 15 topical precision improvement compared with popular clustering techniques.
Graph-Based Approach on Social Data Mining

Abstract:Powered by big data infrastructures, social network platforms are gathering data on many aspects of our daily lives. The online social world is reflecting our physical world in an increasingly detailed way by collecting people's individual biographies and their various of relationships with other people. Although massive amount of social data has been gathered, an urgent challenge remain unsolved, which is to discover meaningful knowledge that can empower the social platforms to really understand their users from different perspectives. Motivated by this trend, my research addresses the reasoning and mathematical modeling behind interesting phenomena on social networks. Proposing graph based data mining framework regarding to heterogeneous data sources is the major goal of my research. The algorithms, by design, utilize graph structure with heterogeneous link and node features to creatively represent social networks' basic structures and phenomena on top of them. The graph based heterogeneous mining methodology is proved to be effective on a series of knowledge discovery topics, including network structure and macro social pattern mining such as magnet community detection~\cite{GuanKDD12}, social influence propagation and social similarity mining~\cite{GuanCIKM12}, and spam detection~\cite{GuanICDM11}. The future work is to consider dynamic relation on social data mining and how graph based approaches adapt from the new situations.

Abstract:How to unearth relationships of network users is a hot spot of social network research fields.In some famous social network websites,such as RenRen.com and Facebook,relationship is characterized by users' registration information,but for users of BBS and micro-blog,the relationship can not characterize by registration information.Therefore,according to features of BBS users,this paper introduced the concept of cognition degree to describe the behavior of users' interactions.Furthermore,it proposed a community relationship mining algorithm based on users' cognition degree.At the same time,it put forward a visual presentation method.This method could intuitively show communities of BBS users and their classifications.Experiments on http://smth.edu.cn and other BBS systems show the method above has a good performance.

Abstract:In recent years, the study of real-world graphs has revealed their inherent heterogeneity, prompting growing research interest in heterogeneous graphs. Characterized by diverse node and relation types, heterogeneous graphs have led to the development of heterogeneous graph neural networks, which possess the remarkable ability of modeling such heterogeneity. Consequently, researchers have embraced these networks, applying them in various domains. A prevalent approach is using meta-path based methods in heterogeneous graph neural networks. However, a significant limitation arises from the fact that such methods tend to overlook vital attribute information within intermediate nodes and disregard relevant semantics across various meta-paths. To address the above limitations, we propose a new model named HGNN-MRCS. Specifically, HGNN-MRCS incorporates three key components, i.e., a relation aware module to encapsulate the attribute information of the intermediate nodes; a meta-path aware technique to facilitate learning of semantic information of each meta-path and enable higher-order representation learning; and a knowledge distillation strategy to learn relevant semantics across meta-paths and fuse them. Experimental results on four real-world datasets demonstrate the superior performance of this work over the SOAT methods. Abstract:Collaborative filtering algorithms haven been widely used in recommender systems. However, they often suffer from the data sparsity and cold start problems. With the increasing popularity of social media, these problems may be solved by using social-based recommendation. Social-based recommendation, as an emerging research area, uses social information to help mitigate the data sparsity and cold start problems, and it has been demonstrated that the social-based recommendation algorithms can efficiently improve the recommendation performance. However, few of the existing algorithms have considered using multiple types of relations within one social network. In this paper, we investigate the social-based recommendation algorithms on heterogeneous social networks and proposed Hete-CF, a Social Collaborative Filtering algorithm using heterogeneous relations. Distinct from the exiting methods, Hete-CF can effectively utilize multiple types of relations in a heterogeneous social network. In addition, Hete-CF is a general approach and can be used in arbitrary social networks, including event based social networks, location based social networks, and any other types of heterogeneous information networks associated with social information. The experimental results on two real-world data sets, DBLP (a typical heterogeneous information network) and Meetup (a typical event based social network) show the effectiveness and efficiency of our algorithm.
