Abstract:Rationally fixing operation optimization target values of thermal power sets is the premise and foundation of effectuating performance evaluation and operation optimization, which is the key for the power station to save energy and reduce consumption. The paper proposes using data mining to find the optimization target value of controllable parameters. Based on the history data stored in supervisory information system of a 600 WM unit, firstly, a clustering method is used to construct fuzzy sets for the steady-state operating data under specific operation condition. Then, fuzzy association rules mining algorithm is used to get the operating target values when the power consumption rate is relatively low. Thus the operation optimization curve can be obtained to guide the practical operation.

Abstract:This paper studies the problem of wide working conditions operational performance optimization of steam turbine units in coal-fired thermal power plants. A method based on big data association rule mining is proposed to establish relationships between a set of key controllable operating parameters and heat consumption rate of the units and then to determine optimal target values of the operating parameters. To deal with sparse data discretized from continuous unit operating data, a new association rule mining algorithm is proposed firstly. It utilizes a binary matrix to store data and introduces a search technique which combines linked list with pointers to mine frequent itemsets. These greatly eliminate the impact of sparsity of data i.e., large differences among transactions and scattered item distribution, on performance of the mining algorithm. Furthermore, in order to process large-scale data efficiently, a parallel implementation of the algorithm on Apache Spark platform is given. Finally, taking a steam turbine in a 600MW subcritical thermal power unit in China as an example, an overall optimization procedure including association rule mining and target value acquiring is presented. The mining results show that the target values calculated by the proposed optimization method can reduce heat consumption rate of the unit and improve economic benefits of the power plant significantly. Note to Practitioners —This research is motivated by the urgent requirement for energy saving and pollutant emission reducing in todays coal-fired power plants, especially in old thermal power plants. To achieve this objective, an effective method is to determine target values (also known as optimal values or benchmark values) of some key controllable operating parameters to realize operating optimization of the thermal power units. Existing target value determination approaches usually adopt the design values or the thermodynamic calculation values, which cannot truly represent the changes of unit operating characteristics. This research proposes a new big data-driven steam turbine unit target value determination method using association rule mining to reduce heat consumption rate of the unit. We not only design a new association rule mining algorithm but also give a parallel implementation of it on advanced big data distributed parallel computing framework Apache Spark, making the proposed optimization method efficiently mine large scale operating data. The proposed operating optimization method is based on the actual operating data of the unit. It has high reliability and good general applicability for different types of coal-fired power units. The optimization experiment on a steam turbine unit in China shows that the obtained target values are valuable for guiding optimization operation of the unit under wide working conditions. In the future, we will consider explicit pollutant emission in the optimization index and address multi-index operating optimization of the steam turbine unit.

Abstract:As the parameters from the thermal power plant DCS (Distributed Control System) data have closely relationships, the association rules data mining is tried to be applied in the determination the optimization values in the thermal power plant. A model is built by the mining tools Clementine 12.0 based on the GRI (generalized rule induction) algorithm. The analysis on the model shows that the values of controllable operating parameters can be determined in order to improve the thermal efficiency by data mining. Thus such method is helpful for the actual operation in the plant.

Abstract:As the development of electric industry, more and more real-time data are sent to database by DAS and DCS and large amounts of data are accumulated. Abundantly valuable knowledge exists in the history data and it is hard to find and summarize them in traditional way. This paper proposes the operation optimization based on data mining in power plant. The basic structure of the operation optimization based on data mining is established and the fuzzy association rule mining is introduced to find the optimization target value from quantitative values of the equipments in power plant industry process. Based on the history data of a 300MW unit, the optimal values of the operating parameters are found out by data mining techniques. The optimal values are provided to the operators to guide the operation online and the excellent performance is achieved in the power plant.

Abstract:The scale of plant data collected in real-time database by DAS and DCS system in power plant is becoming larger and larger. There are abundant and valuable knowledge hidden behind these data. However, the knowledge discovered from these data through artificial analysis is impractical, hence a method utilizes the data mining technology to serve as a facility for process control and optimization of a power plant is proposed. The basic concept and knowledge of data mining is explained at first, then the application of data mining in two aspects, i.e. dynamic process control and supervisory steady state optimization, which are the most important issue of automatic operation of thermal power equipment is expounded. Finally, a system, which integrated the control and optimization module with the knowledge and rule-base obtained from operation database by data mining method, is proposed.

Abstract:In order to explore potential value of explosively growing data in thermal power unit, this paper proposes a big data mining method based on Hadoop-based Spark cluster-computing framework and algorithms. Firstly, positive and negative balance methods are used to accurately obtain actual net coal consumption, and maximum information coefficient method is used to select all parameters related to optimization objectives. Then, Spark-based Mini-Batch K-means algorithm and Elbow method are constructed to divide whole operating modes. After that, all data are discretized and mapped to corresponding intervals by using Spark-based Elbow method and Mini-Batch K-means algorithm. Finally, Spark-based parallel FP-growth algorithm is used to deeply mine the potential relationships and laws. To verify the proposed method, a 350-MW thermal power unit is taken as a study case. The important conclusions are as follows: (1) the proposed Spark-based Mini-Batch K-means algorithm reduces the calculation time by 57.11% compared with Mini-Batch K-means algorithm, and 85.61% calculation time compared with K-means algorithm. The proposed Spark-based FP-growth algorithm reduces computational time by 32.8% compared with FP-growth algorithm. (2) Strong association rules of whole operating modes are mined, and operating optimization guidance schemes for important parameters are obtained. Take operating mode 1 as an example: if the optimal result can be reasonably applied, it can save 2.942 g coal per kilowatt hour. (3) Besides, we have found out some other potential relationships among parameters, which have important reference value for on-site operators to analyze economy of the thermal power unit.

Abstract:A multi-objective optimization based on improved K-means algorithm for thermal power plant operation is proposed in this paper. First, an improved K-means algorithm that aims at updating the method of selecting the clustering number and initial clustering center is applied to divide unit load and coal quality condition. Furthermore, a multi-objective optimization method is developed to realize the balance between the economic indicator and the environmental indicator, thus the corresponding optimal operation parameters of the two performance indicators for each condition can be obtained, which can effectively guide the power station operation. Lastly, taking the historical operation data of a 300MW unit as the experimental object, the simulation results show that the proposed multi-objective optimization based on improved K-means algorithm in this paper is effective and reasonable for the power station operation.

It therefore is vital for optimizing the operation of power plants. Actual states of operation of thermal power units can often not be correctly reflected by optimization target values determined with traditional methods. A way of operation optimization of thermal power units is proposed by applying power electronic technology for making full use of the large amount of historical data stored in power plants. The optimization target of thermal power units operation is found by applying power electronic technology mining algorithm. As a practical example optimal values for all modes of operation of a certain 300MW power set are found which may be used for guiding targets of fossil fired power plants can raise the power set’s efficiency and reduce the emission of contaminants.

Abstract:Thermal power units are frequently operated at a wide range of working conditions due to fast and large-scale penetration of intermittent renewable power. Most existing modelling based thermal power unit operation optimization methods are developed for either full-load working condition or certain static part-load working conditions. A modelling and optimization framework capable of covering the entire range of working conditions of a thermal power unit remains a challenge. In this work, we propose an operation data based approach to process modelling of thermal power units. Mathematical models are firstly developed for key components of a thermal power unit, including pipes, stages of turbines, heat exchangers and pumps, where performance of these components may change under different working conditions. Characteristics of these components are then calibrated using operation data obtained over a certain period covering various working conditions. With the proposed method, both design and off design performances of a thermal power unit can be monitored. A case study is provided, where the proposed method is applied in a 330MW sub-critical thermal power unit in Shanxi, China. Results show that a substantial increase in the thermal efficiency can be achieved after applying the proposed method.

Abstract:Complicated nonlinear relationships exist among many data in the real-time control-process of large power plant.And data-mining technology could find knowledge,analyze parameters and regulate them.This paper ascertained target-value by means of data-mining,which supported energy-loss analysis.The paper introduced relative theory on data mining,studied and applied target-value model of thermal supervised parameters in the way of clustering algorithm.k-means arithmetic was utilized to analyze real-time operating data of thermal units,and mined target values of pressure loss in reheater and exhaust-gas temperature from boiler.The target-value models for main supervised parameters of boiler were received,which was proved to be effective.And the results supply a new idea and effective method for target-value models.

Abstract:Most real-time optimization (RTO) methods in process industries are based on rigorous (mechanistic) models or on some special performance tests. Both methods are difficult to apply due to low model accuracy and high costs in modeling, in computation or in performance tests. In this work, a real-time optimization method based on system identification is developed. No rigorous models or special performance tests are needed in this approach, making it cost-effective and applicable in various process industries and especially suitable for energy and utility systems. First, the selection of objective function and of decision variables is discussed. Then the identification-based optimization method is proposed where a closed-loop multivariable identification approach is incorporated. The method is verified using a simulated power plant and is also partially applied to a real power plant.

Abstract:Desulfurization systems in coal-fired power stations often suffer the problem of high operating costs caused by a rule-of-thumb control strategy, which implies great potential for optimization of the operation. Due to the complex desulfurization mechanism, frequently fluctuating unit load, and severe disturbance, it is challenging to determine the optimal operating parameters based on the traditional mechanistic models, and the operating parameters are closely related to the operational efficiency of the flue gas desulfurization system. In this paper, an operation strategy optimization method for the desulfurization process is proposed based on a data mining framework, which is able to determine online the optimal operating parameter settings from a large amount of historical data. First, Principal Component Analysis (PCA) is used to reduce data redundancy by mapping the data into a new vector space. Based on the new vector space, an enhanced fuzzy C-means clustering (Enhanced-FCM) is developed to cluster the historical data into groups sharing similar characteristics. Taking sulfur dioxide emission concentration as a constraint condition, the system is optimized with economic benefits and desulfurization efficiency as the objective function. When performing optimization, the group that current operating conditions belong to is determined first, then the operating parameters of the best performance are searched within the group and provided as the optimization results. The method is validated and tested based on the data from a wet flue gas desulfurization (WFGD) system of a 1000 MWe supercritical coal-fired power plant in China. The results indicate that the proposed operation strategy can appropriately obtain operating parameter settings at different conditions, and effectively reduce the desulfurization cost under the constraint of meeting emission requirements. Abstract:With the aim of reducing energy con sumption in power plants,the load optimization allocation method of thermal power plants is studied,and a new load allocation method is proposed:By utilizing massive historical data of the unit and combining big data analysis and processing techniques,a case library for unit load optimization and allocation is established.Real time load,coal quality parameters,environmental temperature,and other factors are matched with the case library.TOPSIS is used to establish comprehensive evaluation indicators,and subjective and objective weighting methods are used to combine EWM and AHP to obtain combined weights and provide suggestions for load optimization and allocation.Finally,numerical examples show that the proposed method has fast solving speed and can comprehensively consider subjective and objective factors for multi-objective optimization under the condition of meeting the total load instructions,demonstrating the effectiveness of the proposed method.

Abstract:In the near and medium term, thermal power generation will still play an important peak-shaving role in providing grid connection to volatile renewable energy. Thermal power units need to adjust from the current load to the given load within a given time period, which provides space for operational improvement. In this paper, we propose an operating improvement method for the thermal power unit based on real-time monitoring data by observation dividing, feature construction and selection, clustering, and machine learning. The unit operation data is categorized into three feature subsets based on domain knowledge, which is used to distinguish different functions of historical data. Subsequently, the optimal feature subset and observations are selected for building regression models, including linear regression (LR), ensemble tree regression (ETR), neural network regression (NNR), and support vector regression (SVR). R-squared (R 2 ), root mean square error (RMSE), and mean absolute error (MAE) are adopted to test the performance of the proposed regression model on the real-time monitoring data of a thermal unit, which has 80,000 observations of 36 different variables. Compared with benchmark methods, the proposed method has lower regression error in the numerical experiment. Thus, we can thereby improve the efficiency of operational management based on the built learning model. Furthermore, in response to peak shaving requirements, the proposed method in this article considers operational optimization over time periods containing multiple time points compared to the traditional operational optimization perspective. With the continuous arrival of monitoring data, the above method can be updated in a timely manner based on the new database to address model adjustments caused by unit aging and other factors.

Abstract:The operation optimization of thermal power units is of great significance for energy saving and consumption reduction. Under certain boundary constraints, determining the target value of adjustable parameters is the key to optimal operation of the unit. The basic method is to analyse the historical operation data, from where select the data with the best performance indicators in all range of working condition as the target sample, to establish the model between the boundary parameters and the adjustable parameters. The most difficult step is to solve the conditional probability distribution of the performance parameters with respect to the boundary parameters. In this paper, a hierarchical regression method is proposed to slice the raw data about the performance index, and the historical data is conditionally segmented. Based on this, a modelling framework is designed for the target value of the adjustable parameters of the thermal power unit. Finally, the operation data of an ultra-supercritical 1000MW thermal power unit is selected for verification. The results show that the method has the advantages of stable, and can provide the adjustment direction for the optimal operation of thermal power units.

Abstract:The management of reactive resources plays an important role in maintaining voltage stability and system reliability. This paper presents a new method to find the optimal solution to reactive regulation in power system, using the daily data collected in power substations. The new algorithm is combined with improved ant colony algorithm and Apriori data mining technique. The mathematic models of reactive optimization are described and applied to the reactive optimal compensation in an example electric system. Test results show that the application of the new algorithm proposed in this paper for determining the plan of reactive optimization operation can raise the system’s operation efficiency and reduce the power loss.

Abstract:The present generation of district heating (DH) technologies will have to be further developed into the 4th generation to fulfil the important role in future smart energy systems. At present, automatic meter reading systems have been installed in DH systems. These systems make hourly or even minutely meter readings available at low cost. However, the sheer quantity and complex of the data poses a challenge at various levels for traditional data analysis approaches. Data mining is a promising technology and is used to automatically extract valuable knowledge hidden in large amounts of data. To investigate the potential application of descriptive data mining techniques in DH systems, this study proposes a method based on descriptive data mining to improve the energy performance of DH substations. The proposed method consists of five steps: data cleaning, data transformation, cluster analysis, association analysis, and interpretation/evaluation. Data cleaning and transformation are implemented to improve data quality and transform data into forms that are appropriate for mining. Cluster analysis is performed to identify distinct operating patterns of substations. Based on each pattern, association analysis is then adopted to discover the unsuspected knowledge in the form of rules. Interpretation/ evaluation is performed to select and interpret potentially useful rules. To demonstrate its applicability, the proposed method is used to analyze the datasets obtained from an automatic meter reading system at two substations in the DH system in Changchun, China. This application reveals that the method can effectively extract potentially useful knowledge and thereby provide essential guidance for the fault detection and operation optimization of DH substations.

Abstract:Coal-fired thermal power plants, which represent the largest proportion of China's electric power system, are very sluggish in responding to power system load demands. Thus, a reasonable and feasible scheme for the medium-term optimal commitment of thermal units (MOCTU) can ensure that the generation process runs smoothly and minimizes the start-up and shut-down times of thermal units. In this paper, based on the real-world and practical demands of power dispatch centers in China, a flexible mathematical model for MOCTU that uses equal utilization hours for the installed capacity of all thermal power plants as the optimization goal and that considers the award hours for MOCTU is developed. MOCTU is a unit commitment (UC) problem with characteristics of large-scale, high dimensions and nonlinearity. For optimization, an improved progressive optimality algorithm (IPOA) offering the advantages of POA is adopted to overcome the drawback of POA of easily falling into the local optima. In the optimization process, strategies of system operating capacity equalization and single station operating peak combination are introduced to move the target solution from the boundary constraints along the target isopleths into the feasible solution's interior to guarantee the global optima. The results of a case study consisting of nine thermal power plants with 27 units show that the presented algorithm can obtain an optimal solution and is competent in solving the MOCTU with high efficiency and accuracy as well as that the developed simulation model can be applied to practical engineering needs.

Abstract:Automatic meter reading system is capable of collecting and storing a huge number of district heating (DH) data. However, the data obtained are rarely fully utilized. Data mining is a promising technology to discover potential interesting knowledge from vast data. This paper applies data mining methods to analyse the massive data for improving energy performance of DH substation. The technical approach contains three steps: data selection, cluster analysis and association rule mining (ARM). Two-heating-season data of a substation are used for case study. Cluster analysis identifies six distinct heating patterns based on the primary heat of the substation. ARM reveals that secondary pressure difference and secondary flow rate have a strong correlation. Using the discovered rules, a fault occurring in remote flow meter installed at secondary network is detected accurately. The application demonstrates that data mining techniques can effectively extrapolate potential useful knowledge to better understand substation operation strategies and improve substation energy performance.
