Abstract:Scalable image retrieval systems usually involve hierarchical quantization of local image descriptors, which produces a visual vocabulary for inverted indexing of images. Although hierarchical quantization has the merit of retrieval efficiency, the resulting visual vocabulary representation usually faces two crucial problems: (1) hierarchical quantization errors and biases in the generation of "visual words"; (2) the model cannot adapt to database variance. In this paper, we describe an unsupervised optimization strategy in generating the hierarchy structure of visual vocabulary, which produces a more effective and adaptive retrieval model for large-scale search. We adopt a novel Density-based Metric Learning (DML) algorithm, which corrects word quantization bias without supervision in hierarchy optimization, based on which we present a hierarchical rejection chain for efficient online search based on the vocabulary hierarchy. We also discovered that by hierarchy optimization, efficient and effective transfer of a retrieval model across different databases is feasible. We deployed a large-scale image retrieval system using a vocabulary tree model to validate our advances. Experiments on UKBench and street-side urban scene databases demonstrated the effectiveness of our hierarchy optimization approach in comparison with state-of-the-art methods.
Large-scale Image Retrieval Based on Boosting Iterative Quantization Hashing with Query-Adaptive Reranking.

Abstract:Image hashing based Approximate Nearest Neighbor (ANN) searching has drawn more and more attention in large-scale image dataset applications. It is still challenging to learn hashing codes to achieve good search performance. In this paper, we propose an image retrieval method based on boosting iterative quantization hashing method with query-adaptive reranking. Firstly, in boosting iterative quantization hashing embedding, we adopt boosting-based method to generate inputs to learn hashing functions. Then we optimize the hashing functions with a loss function by considering the relationship between samples. Once the hashing codes are generated, Query-Adaptive Reranking (QAR) method is proposed to learn bit-level weights for each category and query-adaptive weights for each hashing bit. In this way, the discrete Hamming distance value can be continuous, and many irrelevant returned images can be sorted to the back. We conduct experiments on three public datasets, and comparison results with six state-of-the-art methods to illustrate the effectiveness of the proposed method.
Nonlinear Discrete Cross-Modal Hashing for Visual-Textual Data

Abstract:Hashing techniques have been widely adopted for cross-modal retrieval due to their low storage cost and fast query speed. Recently, some unimodal hashing methods have tried to directly optimize the objective function with discrete binary constraints. Inspired by these methods, the authors propose a novel supervised cross-modal hashing method called Discrete Cross-Modal Hashing (DCMH) to learn the binary codes without relaxing them. DCMH is formulated through semantic similarity reconstruction, and it learns binary codes for use as ideal features for classification. Furthermore, DCMH alternately updates binary codes for each modality, and its discrete hashing codes are learned efficiently, bit by bit, which is quite promising for large-scale datasets. To evaluate the effectiveness of the proposed discrete optimization, the authors optimize their objective function in a relax-and-threshold manner. Extensive empirical results on both image-text and image-tag datasets demonstrate that DCMH is a significant improvement over previous approaches in terms of training time and retrieval performance.

Abstract:Supervised cross-modal hashing has gained increasing research interest on large-scale retrieval task owning to its satisfactory performance and efficiency. However, there are still some issues to be further addressed: (1) most of them fail to capture the inherent data structure effectively due to the complex correlations among heterogeneous data points; (2) most of them obtain continuous solutions firstly and then quantize the continuous solutions to generate hash codes directly, which causes large quantization error and consequent suboptimal retrieval performance; (3) most of them suffer from relatively high memory cost and computational complexity during training procedure, which makes them unscalable. In this paper, to address above issues, we propose a supervised hashing method for cross-modal retrieval dubbed Efficient Discrete Supervised Hashing (EDSH). Specifically, the sharing space learning with collective matrix factorization and semantic embedding with class labels are seamlessly integrated to learn hash codes. Therefore, the feature based similarities and semantic correlations are both preserved in hash codes, which makes the learned hash codes more discriminative. Then an efficient discrete optimal scheme is designed to handle the scalable issue. Instead of learning hash codes bit-by-bit, hash codes matrix can be obtained directly which is more efficient. Extensive experimental results on three public datasets show that our EDSH produces a superior performance in both accuracy and scalability over several existing cross-modal hashing approaches.

Abstract:In this paper, we focus on the hierarchy and discriminating ability of visual vocabulary.We propose to use the category information of images and the spatial context of keypoints to select appropriate visual words from different hierarchical levels.Existing approaches, such as flat vocabulary and vocabulary tree, can change the hierarchy of all visual words at the same time, by setting different cluster numbers and tree height respectively.However, the most appropriate visual words may be at different hierarchical levels, and existing approaches could not adjust the hierarchy of different visual words separately.To address this problem, we propose an object function to describe the consistence of visual words, with category information of images and spatial context of keypoints, and then we adopt simulated annealing algorithm to search for a sub-optimal solution, which corresponds to a visual vocabulary selected from the vocabulary tree.Different from existing methods, the proposed approach can select the most appropriate visual words from different levels adaptively, which can improve the performances in image annotation and classification tasks.Experiments on widely-used 15-scenes dataset demonstrate the effectiveness of the proposed approach.
Learning to Distribute Vocabulary Indexing for Scalable Visual Search

Abstract:In recent years, there is an ever-increasing research focus on Bag-of-Words based near duplicate visual search paradigm with inverted indexing. One fundamental yet unexploited challenge is how to maintain the large indexing structures within a single server subject to its memory constraint, which is extremely hard to scale up to millions or even billions of images. In this paper, we propose to parallelize the near duplicate visual search architecture to index millions of images over multiple servers, including the distribution of both visual vocabulary and the corresponding indexing structure. We optimize the distribution of vocabulary indexing from a machine learning perspective, which provides a “memory light” search paradigm that leverages the computational power across multiple servers to reduce the search latency. Especially, our solution addresses two essential issues: “What to distribute” and “How to distribute”. “What to distribute” is addressed by a “lossy” vocabulary Boosting, which discards both frequent and indiscriminating words prior to distribution. “How to distribute” is addressed by learning an optimal distribution function, which maximizes the uniformity of assigning the words of a given query to multiple servers. We validate the distributed vocabulary indexing scheme in a real world location search system over 10 million landmark images. Comparing to the state-of-the-art alternatives of single-server search , , and distributed search , our scheme has yielded a significant gain of about 200% speedup at comparable precision by distributing only 5% words. We also report excellent robustness even when partial servers crash.

Abstract:This work aims at developing a scalable vision-based location recognition system where the backend database can be updated incrementally. Our proposed framework enables incremental indexing of vocabulary tree model, which efficiently includes new data into model refinement without re-generating entire model from overall dataset. An adaption trigger criterion is presented to lessen system computational cost, which is achieved by density-based relative entropy estimation between original dataset and newly coming data. Experiments on Seattle urban scene datasets with over 20 K street-side images show the effectiveness of our work.

Abstract:Constructing discriminative feature descriptors is crucial towards effective image retrieval. The state-of-the-art powerful global descriptor for this purpose is Vector of Locally Aggregated Descriptors (VLAD). Given a set of local features (say, SIFT) extracted from an image, the VLAD is generated by quantizing local features with a small visual vocabulary (64 to 512 centroids), aggregating the residual statistics of quantized features for each centroid and concatenating the aggregated residual vectors from each centroid. One can increase the search accuracy by increasing the size of vocabulary (from hundreds to hundreds of thousands), which, however, it leads to heavy computation cost with flat quantization. In this paper, we propose a hierarchical multi-VLAD to seek the tradeoff between descriptor discriminability and computation complexity. We build up a tree-structured hierarchical quantization (TSHQ) to accelerate the VLAD computation with a large vocabulary. As quantization error may propagate from root to leaf node (centroid) with TSHQ, we introduce multi-VLAD, which constructing a VLAD descriptor for each level of the vocabulary tree, so as to compensate for the quantization error at that level. Extensive evaluation over benchmark datasets has shown that the proposed approach outperforms state-of-the-art in terms of retrieval accuracy, fast extraction, as well as light memory cost.

Abstract:Bag-of-Words (BoW) model based on SIFT has been widely used in large scale image retrieval applications. Feature quantization plays a crucial role in BoW model, which generates visual words from the high dimensional SIFT features, so as to adapt to the inverted file structure for indexing. Traditional feature quantization approaches suffer several problems: 1) high computational cost---visual words generation (codebook construction) is time consuming especially with large amount of features; 2) limited reliability---different collections of images may produce totally different codebooks and quantization error is hard to be controlled; 3) update inefficiency--once the codebook is constructed, it is not easy to be updated. In this paper, a novel feature quantization algorithm, scalar quantization , is proposed. With scalar quantization, a SIFT feature is quantized to a descriptive and discriminative bit-vector, of which the first tens of bits are taken out as code word . Our quantizer is independent of collections of images. In addition, the result of scalar quantization naturally lends itself to adapt to the classic inverted file structure for image indexing. Moreover, the quantization error can be flexibly reduced and controlled by efficiently enumerating nearest neighbors of code words. The performance of scalar quantization has been evaluated in partial-duplicate Web image search on a database of one million images. Experiments reveal that the proposed scalar quantization achieves a relatively 42% improvement in mean average precision over the baseline (hierarchical visual vocabulary tree approach), and also outperforms the state-of-the-art Hamming Embedding approach and soft assignment method.

Abstract:Object retrieval in the large-scale image corpus is an appealing, yet challenging task. Most of existing frameworks are based on bag-of-visual-words (BoVW) model. However, BoVW has an obvious drawback, i.e. lack of spatial information. In this paper, we propose weighted transformable spatial pyramid and scalable query for object retrieval. We first break the whole image into sub-images and then make these sub-images up in a new order in the final representation. Our method has two contributions: 1) relative spatial relationships of local features instead of absolute geometric layouts of features are encoded so that translation invariance is guaranteed, 2) scaling invariance in the image representation is ensured by scalable query. The experimental results show that our approach outperforms BoVW and traditional spatial pyramid matching.
Large scale partial-duplicate image retrieval with bi-space quantization and geometric consistency

Abstract:The state-of-the-art image retrieval approaches represent image with a high dimensional vector of visual words by quantizing local features, such as SIFT, solely in descriptor space. The resulting visual words usually suffer from the dilemma of discrimination and ambiguity. Besides, geometric relationships among visual words are usually ignored or only used for post-processing such as re-ranking. In this paper, to improve the discriminative power and reduce the ambiguity of visual word, we propose a novel bispace quantization strategy. Local features are quantized to visual words first in descriptor space and then in orientation space. Moreover, geometric consistency constraints are embedded into the relevance formulation. Experiments in web image search with a database of one million images show that our approach achieves an improvement of 65.4% over the baseline bag-of-words approach.

Abstract:Hashing has been widely applied to approximate nearest neighbor search for large-scale multimedia retrieval. Supervised hashing improves the quality of hash coding by exploiting the semantic similarity on data pairs and has received increasing attention recently. For most existing supervised hashing methods for image retrieval, an image is first represented as a vector of hand-crafted or machine-learned features, then quantized by a separate quantization step that generates binary codes. However, suboptimal hash coding may be produced, since the quantization error is not statistically minimized and the feature representation is not optimally compatible with the hash coding. In this paper, we propose a novel Deep Quantization Network (DQN) architecture for supervised hashing, which learns image representation for hash coding and formally control the quantization error. The DQN model constitutes four key components: (1) a sub-network with multiple convolution-pooling layers to capture deep image representations; (2) a fully connected bottleneck layer to generate dimension-reduced representation optimal for hash coding; (3) a pairwise cosine loss layer for similarity-preserving learning; and (4) a product quantization loss for controlling hashing quality and the quantizability of bottleneck representation. Extensive experiments on standard image retrieval datasets show the proposed DQN model yields substantial boosts over latest state-of-the-art hashing methods.
Bayes Merging of Multiple Vocabularies for Scalable Image Retrieval

Abstract:The Bag-of-Words (BoW) representation is well applied to recent state-of-the-art image retrieval works. Typically, multiple vocabularies are generated to correct quantization artifacts and improve recall. However, this routine is corrupted by vocabulary correlation, i.e., overlapping among different vocabularies. Vocabulary correlation leads to an over-counting of the indexed features in the overlapped area, or the intersection set, thus compromising the retrieval accuracy. In order to address the correlation problem while preserve the benefit of high recall, this paper proposes a Bayes merging approach to down-weight the indexed features in the intersection set. Through explicitly modeling the correlation problem in a probabilistic view, a joint similarity on both image- and feature-level is estimated for the indexed features in the intersection set. We evaluate our method through extensive experiments on three benchmark datasets. Albeit simple, Bayes merging can be well applied in various merging tasks, and consistently improves the baselines on multi-vocabulary merging. Moreover, Bayes merging is efficient in terms of both time and memory cost, and yields competitive performance compared with the state-of-the-art methods.

Abstract:Scalable vocabulary tree (SVT) is a data compression structure which gains scalable visual vocabularies from hierarchical k-means clustering of local image features. Due to both high robustness in data retrieval and great potentials to process huge data, it has become one of the state-of-the-art methods building on the bag-of-features. However, such bag-of-words representations mainly suffer from two limitations. The paper gives a performance research of re-ranking in sub-image retrieval using SVT which is built from local Speed Up Robust Features descriptors. Firstly, the paper gives a study on retrieval performance using different single layers of the tree, which tells it divides data too coarsely for low layers with a small quantity of leaf nodes, while too finely for the 6-th layer with too many leaf nodes. Then using the best selected layer, the authors give a comparative analysis with popular advanced re-ranking strategies in the existing literatures. Finally, the authors propose a weighted score method that calculates matching score from dominating layers. The experimental results prove that the weighted score method achieves almost optimal retrieval performance when using SVT for data representations. Meanwhile, it almost doesn’t increase any computational complexity, and can be implemented easily.
Visual Vocabulary Optimization with Spatial Context for Image Annotation and Classification

Abstract:In this paper, we propose a new approach of visual vocabulary optimization with spatial context, which contains important spatial information that has not been fully exploited. The novelty of our method mainly lies in two aspects: when spatial information is considered, and how spatial information is used. For the first aspect, the existing methods generally consider spatial information after the visual vocabulary is built, while we employ the spatial information in the construction of visual vocabulary, to produce more accurate visual vocabulary. For the second aspect, different from existing methods which use spatial information to re-rank the original retrieval results, to generate the local keypoint groups such as visual phrases, or in spatial pyramid matching kernel, etc, we propose a novel method that employs spatial information as side information to constrain the construction of visual vocabulary. Instead of simply assigning keypoints to the nearest cluster centers, we also take the spatial context of keypoints into consideration in the clustering process. With the proposed approach, more accurate visual vocabulary can be generated, and the evaluation results can be improved in both image annotation and classification tasks. Experiments on widely-used 15-scenes dataset demonstrate the effectiveness of the proposed approach.
Sub-Selective Quantization for Large-Scale Image Search

Abstract:Recently with the explosive growth of visual content on the Internet, large-scale image search has attracted intensive attention. It has been shown that mapping highdimensional image descriptors to compact binary codes can lead to considerable efficiency gains in both storage and similarity computation of images. However, most existing methods still suffer from expensive training devoted to large-scale binary code learning. To address this issue, we propose a sub-selection based matrix manipulation algorithm which can significantly reduce the computational cost of code learning. As case studies, we apply the sub-selection algorithm to two popular quantization techniques PCA Quantization (PCAQ) and Iterative Quantization (ITQ). Crucially, we can justify the resulting sub-selective quantization by proving its theoretic properties. Extensive experiments are carried out on three image benchmarks with up to one million samples, corroborating the efficacy of the sub-selective quantization method in terms of image retrieval.

Abstract:Deep hashing approaches, including deep quantization and deep binary hashing, have become a common solution to large-scale image retrieval due to their high computation and storage efficiency. Most existing hashing methods cannot produce satisfactory results for fine-grained retrieval, because they usually adopt the outputs of the last CNN layer to generate binary codes. Since deeper layers tend to summarize visual clues, e.g. , texture, into abstract semantics, e.g. , dogs and cats, the feature produced by the last CNN layer is less effective in capturing subtle but discriminative visual details that mostly exist in shallow layers. To improve fine-grained image hashing, we propose P yramid H ybrid P ooling Q uantization ( PHPQ ). Specifically, we propose a P yramid H ybrid P ooling ( PHP ) module to capture and preserve fine-grained semantic information from multi-level features, which emphasizes the subtle discrimination of different sub-categories. Besides, we propose a learnable quantization module with a partial codebook attention mechanism , which helps to optimize the most relevant codewords and improves the quantization. Comprehensive experiments on two widely-used public benchmarks, i.e. , CUB-200-2011 and Stanford Dogs, demonstrate that PHPQ outperforms state-of-the-art methods.

Abstract:Hashing has been widely used in large-scale image retrieval based on approximate nearest neighbor search. Most learning-to-hashing methods adopt a two-stage algorithm to generate binary codes. First, original images are mapped into continuous visual features. Then, binary codes are generated by quantization step or separate projection. Nevertheless, these methods are sensitive to quantization operation, i.e., thresholding. To explicitly address this issue, this study proposes a novel feature quantization scheme with a loopy recurrent neural network, called loopy residual hashing, for the purpose of high accuracy in image retrieval. Instead of one-off thresholding-based feature binarization, the proposed approach performs an iterative threshold-then-approximate operation, which calculates the quantization residual after each thresholding step and then imitates another round of binarization to further approximate the coding residual. The resulting sequences of binary codes possess higher representation accuracy and extensive experiments on image retrieval demonstrate its superior discriminative capability over the prior art. In the meantime, theoretical approximation error analysis is given.
Personalized Visual Vocabulary Adaption for Social Image Retrieval

Abstract:With the popularity of mobile devices and social networks, users can easily build their personalized image sets. Thus, personalized image analysis, indexing, and retrieval have become important topics in social media analysis. Because of users' diverse preferences, their personalized image sets are usually related to specific topics and show large feature distribution bias from general Internet images. Therefore, the visual vocabulary trained on general Internet images may could not fit across users' personalized image sets very well. To improve the image retrieval performance on personalized image sets, we propose the personalized visual vocabulary adaption which removes non-discriminative visual words and replaces them with more exact and discriminative ones, i.e., adapt a general vocabulary toward a specific user's image set. The proposed algorithm updates the visual vocabulary during off-line feature quantization, and operates on a limited number of visual words, hence shows satisfying efficiency. Extensive experiments of image search on public datasets demonstrate the efficiency and superior performance of our approach.
