Convergence of Relativistic GANs With Zero-Centered Gradient Penalties

Abstract:Generative adversarial networks (GANs) are prone to mode collapse and non-convergence issues. Relativistic GANs (RpGANs) have been proposed as an alternative to combat mode collapse, but their convergence behavior remains unexplored. In this paper, we use a toy example to demonstrate that unregularized RpGANs do not converge in general. We then introduce zero-centered gradient penalties to address this issue and establish that regularized RpGANs enjoy the same guarantee of local convergence as the original GANs with zero-centered gradient penalties. We further evaluate the effectiveness of gradient-penalized RpGANs on StackedMNIST, where the model achieves full mode coverage and the smallest KL divergence, while maintaining superior stability throughout the course of training. Overall, our re-sults demonstrate that gradient-penalized RpGANs offer a solution to both mode collapse and non-convergence issues in GANs.
