Abstract:Techniques to predict participants’ personality traits in real-time are not yet developed or well-studied. The objective of the current study was to explore the use of gaze and behavioral metrics and machine learning techniques in a hybrid foraging search task to infer an individual's personality traits to enable personalized interaction. We recruited and collected data from 40 university student participants in a hybrid foraging search task experiment. Specifically, the metrics were extracted from different time window sizes (5s, 10s, 15s, and 20s), which referred to the length of time before the participant stopped searching the current screen. Hierarchical clustering analysis was performed on the personality traits scores to group the participants into three groups, namely neuroticism (47.50%), conscientiousness (25.00%), and agreeableness (27.50%). Machine learning models were trained using the eye-gaze and behavioral metrics as inputs and personality trait groups as labels using well-known algorithms (including random forest (RF), support vector machine (SVM), k- nearest neighbor (kNN), and artificial neural network (ANN)). The results from the machine learning modeling showed that the prediction accuracy increased as the window size increased in general. The highest prediction accuracy (83%) was achieved with the kNN algorithm with a 15s time window. Combining eye-gaze and behavioral metrics as input features usually resulted in a better-performing model compared to using eye-gaze metrics alone (up to 10% improvement in accuracy). The current results can be to implement this approach in a brief game-like activity to infer a user's personality traits to enable subsequent intelligent user interface adaptations.

Abstract:Introduction: Personality plays a crucial role in shaping an individual's interactions with the world. The Big Five personality traits are widely used frameworks that help describe people's psychological behaviours. These traits predict how individuals behave within an organizational setting. Methods: In this article, we introduce a virtual reality (VR) strategy for relatively scoring an individual's personality to evaluate the feasibility of predicting personality traits from implicit measures captured from users interacting in VR simulations of different organizational situations. Specifically, eye-tracking and decision-making patterns were used to classify individuals according to their level in each of the Big Five dimensions using statistical machine learning (ML) methods. The virtual environment was designed using an evidence-centered design approach. Results: The dimensions were assessed using NEO-FFI inventory. A random forest ML model provided 83% accuracy in predicting agreeableness. A k -nearest neighbour ML model provided 75%, 75%, and 77% accuracy in predicting openness, neuroticism, and conscientiousness, respectively. A support vector machine model provided 85% accuracy for predicting extraversion. These analyses indicated that the dimensions could be differentiated by eye-gaze patterns and behaviours during immersive VR. Discussion: Eye-tracking measures contributed more significantly to this differentiation than the behavioural metrics. Currently, we have obtained promising results with our group of participants, but to ensure the robustness and generalizability of our findings, it is imperative to replicate the study with a considerably larger sample. This study demonstrates the potential of VR and ML to recognize personality traits.

Gaze-based Human Intention Prediction in the Hybrid Foraging Search Task

Abstract:An agent’s ability to predict a human’s intention can facilitate the effectiveness of a human-agent team. The aim of this study was to explore the feasibility of predicting human intention in the hybrid foraging search task using eye gaze data and machine learning. In the hybrid foraging search paradigm, the human performs searches in patches and decides to stay and exploit a patch or to leave and explore another patch. Researchers have modeled the “patch-leaving problem” on the collective level using the marginal value theorem. However, few have attempted to predict the exact moment when the human will leave. In the current study, 40 participants performed the hybrid foraging search task while eye gaze data were collected with an eye-tracker. The leaving intention was associated with larger pupil size, shorter average fixation duration, larger number of fixations, longer saccade amplitude, and faster saccade velocity compared to the searching intention. A cross-subject machine learning model with an artificial neural network algorithm was able to predict whether a participant would leave the current patch with up to 78% accuracy with a 2-second data analysis window. The length of the data analysis window did not significantly affect prediction accuracy. Furthermore, the earlier the behavior prediction was made, the lower the reliability of the prediction. These results demonstrate that eye gaze features and machine learning algorithms are useful in predicting human intention in visual search tasks.

Abstract:Understanding human visual attention in immersive virtual reality (VR) is crucial for many important applications, including gaze prediction, gaze guidance, and gaze-contingent rendering. However, previous works on visual attention analysis typically only explored one specific VR task and paid less attention to the differences between different tasks. Moreover, existing task recognition methods typically focused on 2D viewing conditions and only explored the effectiveness of human eye movements. We first collect eye and head movements of 30 participants performing four tasks, i.e., Free viewing, Visual search, Saliency, and Track, in 15 360-degree VR videos. Using this dataset, we analyze the patterns of human eye and head movements and reveal significant differences across different tasks in terms of fixation duration, saccade amplitude, head rotation velocity, and eye-head coordination. We then propose EHTask - a novel learning-based method that employs eye and head movements to recognize user tasks in VR. We show that our method significantly outperforms the state-of-the-art methods derived from 2D viewing conditions both on our dataset (accuracy of 84.4% versus 62.8%) and on a real-world dataset ( 61.9% versus 44.1%). As such, our work provides meaningful insights into human visual attention under different VR tasks and guides future work on recognizing user tasks in VR.

Abstract:Virtual reality (VR) is not a new technology but has been in development for decades, driven by advances in computer technology. Currently, VR technology is increasingly being used in applications to enable immersive, yet controlled research settings. Education and entertainment are two important application areas, where VR has been considered a key enabler of immersive experiences and their further advancement. At the same time, the study of human behavior in such innovative environments is expected to contribute to a better design of VR applications. Therefore, modern VR devices are consistently equipped with eye-tracking technology, enabling thus further studies of human behavior through the collection of process data. In particular, eye-tracking technology in combination with machine learning techniques and explainable models can provide new insights for a deeper understanding of human behavior during immersion in virtual environments. In this work, a systematic computational framework based on eye-tracking and behavioral user data and state-of-the-art machine learning approaches is proposed to understand human behavior and individual differences in VR contexts. This computational framework is then employed in three user studies across two different domains. In the educational domain, two different immersive VR classrooms were created where students can learn and teachers can train. In terms of VR entertainment, eye movements open a new avenue to evaluate VR locomotion techniques from the perspective of user cognitive load and user experience. This work paves the way for assessing human behavior in VR scenarios and provides profound insights into the way of designing, evaluating, and improving interactive VR systems. In particular, more effective and customizable virtual environments can be created to provide users with tailored experiences.
Stronger reactivity to social gaze in virtual reality compared to a classical laboratory environment

Abstract:People show a robust tendency to gaze at other human beings when viewing images or videos, but were also found to relatively avoid gaze at others in several real-world situations. This discrepancy, along with theoretical considerations, spawned doubts about the appropriateness of classical laboratory-based experimental paradigms in social attention research. Several researchers instead suggested the use of immersive virtual scenarios in eliciting and measuring naturalistic attentional patterns, but the field, struggling with methodological challenges, still needs to establish the advantages of this approach. Here, we show using eye-tracking in a complex social scenario displayed in virtual reality that participants show enhanced attention towards the face of an avatar at near distance and demonstrate an increased reactivity towards her social gaze as compared to participants who viewed the same scene on a computer monitor. The present study suggests that reactive virtual agents observed in immersive virtual reality can elicit natural modes of information processing and can help to conduct ecologically more valid experiments while maintaining high experimental control.

Abstract:Human visual attention in immersive virtual reality (VR) is key for many important applications, such as content design, gaze-contingent rendering, or gaze-based interaction. However, prior works typically focused on free-viewing conditions that have limited relevance for practical applications. We first collect eye tracking data of 27 participants performing a visual search task in four immersive VR environments. Based on this dataset, we provide a comprehensive analysis of the collected data and reveal correlations between users' eye fixations and other factors, i.e. users' historical gaze positions, task-related objects, saliency information of the VR content, and users' head rotation velocities. Based on this analysis, we propose FixationNet - a novel learning-based model to forecast users' eye fixations in the near future in VR. We evaluate the performance of our model for free-viewing and task-oriented settings and show that it outperforms the state of the art by a large margin of 19.8% (from a mean error of 2.93° to 2.35°) in free-viewing and of 15.1% (from 2.05° to 1.74°) in task-oriented situations. As such, our work provides new insights into task-oriented attention in virtual environments and guides future work on this important topic in VR research.

Abstract:Background: Eye tracking technology is receiving increased attention in the field of virtual reality. Specifically, future gaze prediction is crucial in pre-computation for many applications such as gaze-contingent rendering, advertisement placement, and content-based design. To explore future gaze prediction, it is necessary to analyze the temporal continuity of visual attention in immersive virtual reality. Methods: In this paper, the concept of temporal continuity of visual attention is presented. Subsequently, an autocorrelation function method is proposed to evaluate the temporal continuity. Thereafter, the temporal continuity is analyzed in both free-viewing and task-oriented conditions. Results: Specifically, in free-viewing conditions, the analysis of a free-viewing gaze dataset indicates that the temporal continuity performs well only within a short time interval. A task-oriented game scene condition was created and conducted to collect users' gaze data. An analysis of the collected gaze data finds the temporal continuity has a similar performance with that of the free-viewing conditions. Temporal continuity can be applied to future gaze prediction and if it is good, users' current gaze positions can be directly utilized to predict their gaze positions in the future. Conclusions: The current gaze's future prediction performances are further evaluated in both free-viewing and task-oriented conditions and discover that the current gaze can be efficiently applied to the task of short-term future gaze prediction. The task of long-term gaze prediction still remains to be explored.

Abstract:Virtual reality (VR) is a useful tool to study consumer behavior while they are immersed in a realistic scenario. Among several other factors, personality traits have been shown to have a substantial influence on purchasing behavior. The primary objective of this study was to classify consumers based on the Big Five personality domains using their behavior while performing different tasks in a virtual shop. The personality recognition was ascertained using behavioral measures received from VR hardware, including eye-tracking, navigation, posture and interaction. Responses from 60 participants were collected while performing free and directed search tasks in a virtual hypermarket. A set of behavioral features was processed, and the personality domains were recognized using a statistical supervised machine learning classifier algorithm via a support vector machine. The results suggest that the open-mindedness personality type can be classified using eye gaze patterns, while extraversion is related to posture and interactions. However, a combination of signals must be exhibited to detect conscientiousness and negative emotionality. The combination of all measures and tasks provides better classification accuracy for all personality domains. The study indicates that a consumer’s personality can be recognized using the behavioral sensors included in commercial VR devices during a purchase in a virtual retail store.

Abstract:With the proliferation of consumer virtual reality (VR) headsets and creative tools, content creators have started to experiment with new forms of interactive audience experience using immersive media. Understanding user attention and behaviours in virtual environment can greatly inform creative processes in VR. We developed an abstract VR painting and an experimentation system to study audience encounters through eye gaze and movement tracking. The data from a user experiment with 35 participants reveal a range of user activity patterns in art exploration. Deep learning models are used to study the connections between behavioural data and audience background. New integrated methods to visualise user attention as part of the artwork are also developed as a feedback loop to the content creator.

Imperceptible Gaze Guidance Through Ocularity in Virtual Reality

Abstract:We introduce to VR a novel imperceptible gaze guidance technique from a recent discovery that human gaze can be attracted to a cue that contrasts from the background in its perceptually non-distinctive ocularity, defined as the relative difference between inputs to the two eyes. This cue pops out in the saliency map in the primary visual cortex without being overtly visible. We tested this method in an odd-one-out visual search task using eye tracking with 15 participants in VR. When the target was rendered as an ocularity singleton, participants' gaze was drawn to the target faster. Conversely, when a background object served as the ocularity singleton, it distracted gaze from the target. Since ocularity is nearly imperceptible, our method maintains user immersion while guiding attention without noticeable scene alterations and can render object's depth in 3D scenes, creating new possibilities for immersive user experience across diverse VR applications.

Abstract:Speed and consistency of target-shifting play a crucial role in human ability to perform complex tasks. Shifting our gaze between objects of interest quickly and consistently requires changes both in depth and direction. Gaze changes in depth are driven by slow, inconsistent vergence movements which rotate the eyes in opposite directions, while changes in direction are driven by ballistic, consistent movements called saccades, which rotate the eyes in the same direction. In the natural world, most of our eye movements are a combination of both types. While scientific consensus on the nature of saccades exists, vergence and combined movements remain less understood and agreed upon. We eschew the lack of scientific consensus in favor of proposing an operationalized computational model which predicts the speed of any type of gaze movement during target-shifting in 3D. To this end, we conduct a psychophysical study in a stereo VR environment to collect more than 12,000 gaze movement trials, analyze the temporal distribution of the observed gaze movements, and fit a probabilistic model to the data. We perform a series of objective measurements and user studies to validate the model. The results demonstrate its predictive accuracy, generalization, as well as applications for optimizing visual performance by altering content placement. Lastly, we leverage the model to measure differences in human target-changing time relative to the natural world, as well as suggest scene-aware projection depth. By incorporating the complexities and randomness of human oculomotor control, we hope this research will support new behavior-aware metrics for VR/AR display design, interface layout, and gaze-contingent rendering.

PersonalityScanner: Exploring the Validity of Personality Assessment Based on Multimodal Signals in Virtual Reality

Abstract:Human cognition significantly influences expressed behavior and is intrinsically tied to authentic personality traits. Personality assessment plays a pivotal role in various fields, including psychology, education, social media, etc. However, traditional self-report questionnaires can only provide data based on what individuals are willing and able to disclose, thereby lacking objective. Moreover, automated measurements and peer assessments demand significant human effort and resources. In this paper, given the advantages of the Virtual Reality (VR) technique, we develop a VR simulator -- PersonalityScanner, to stimulate cognitive processes and simulate daily behaviors based on an immersive and interactive simulation environment, in which participants carry out a battery of engaging tasks that formulate a natural story of first-day at work. Through this simulator, we collect a synchronous multi-modal dataset with ten modalities, including first/third-person video, audio, text, eye tracking, facial microexpression, pose, depth data, log, and inertial measurement unit. By systematically examining the contributions of different modalities on revealing personality, we demonstrate the superior performance and effectiveness of PersonalityScanner.

This project focuses on a novel energy efficient technique called adiabatic logic which is based on energy recovery principle and power is compared by designing a multiplier. CMOS technology plays a dominant role in designing low power consuming devices, compared to different logic family CMOS has less power dissipation. Adiabatic logic style is said to be an attractive solution for low power electronic applications. By using Adiabatic techniques energy dissipation in PMOS network can be minimized and some of energy stored at load capacitance can be recycled instead of dissipated as heat. Tanner EDA tools are used for simulation.
GazeIntent: Adapting dwell-time selection in VR interaction with real-time intent modeling

Abstract:The use of ML models to predict a user's cognitive state from behavioral data has been studied for various applications which includes predicting the intent to perform selections in VR. We developed a novel technique that uses gaze-based intent models to adapt dwell-time thresholds to aid gaze-only selection. A dataset of users performing selection in arithmetic tasks was used to develop intent prediction models (F1 = 0.94). We developed GazeIntent to adapt selection dwell times based on intent model outputs and conducted an end-user study with returning and new users performing additional tasks with varied selection frequencies. Personalized models for returning users effectively accounted for prior experience and were preferred by 63% of users. Our work provides the field with methods to adapt dwell-based selection to users, account for experience over time, and consider tasks that vary by selection frequency

Abstract:We examined theories of cross-cultural differences in cognitive style on a sample of 242 participants representing five cultural groups (Czechia, Ghana, eastern and western Turkey, and Taiwan). The experiment involved immersive virtual environments consisting of two salient focal objects and a complex background as stimuli, which were presented using virtual reality headsets with integrated eye-tracking devices. The oculomotor patterns confirmed previous general conclusions that Eastern cultures have a more holistic cognitive style, while Western cultures predominantly have an analytic cognitive style. The differences were particularly noticeable between Taiwan and the other samples. However, we found that the broader cultural background of each group was perhaps just as important as geographical location or national boundaries. For example, observed differences between Eastern (more holistic style) and Western Turkey (more analytic style), suggest the possible influence of varying historical and cultural characteristics on the cognitive processing of complex visual stimuli.

Abstract:<italic>Objective:</italic> Mixed-Reality (XR) technologies promise a user experience (UX) that rivals the interactive experience with the real-world. The key facilitators in the design of such a natural UX are that the interaction has zero lag and that users experience no excess mental load. This is difficult to achieve due to technical constraints such as motion-to-photon latency as well as false-positives during gesture-based interaction. <italic>Methods:</italic> In this paper, we explored the use of physiological features to model the user's intent to interact with a virtual reality (VR) environment. Accurate predictions about when users want to express an interaction intent could overcome the limitations of an interactive device that lags behind the intention of a user. The features leveraged in our classification scheme have a low computational cost and are especially useful for fast decoding of users’ mental states. Our work is a further step towards a useful classification of users’ intent to interact, as a high temporal resolution and speed of detection is crucial. This facilitates natural experiences through zero-lag adaptive interfaces.

Capturing Initial Gaze Attraction in Branded Spaces Through VR Eye-Tracking Technology

Abstract:This paper leverages recent strides in virtual reality (VR) technology to dissect user gaze patterns and initial responses in a VR-based in-store environment, with a focus on how visual elements impact attention in Human–Computer Interaction (HCI). Specifically, this exploratory study focuses on brand-centric components such as logos and colors, while also considering individual variables such as gender and design background. Employing a mixed-methods approach, the research combines qualitative and quantitative tools. A VR-integrated eye-tracking system records how participants' gaze behaves in a virtual retail environment. The study collects data from 50 participants in four scenarios: a control store (Case 1), introduction of the brand's logo signage (Case 2), infusion of the brand's primary color (Case 3), and a fusion of logo and color (Case 4). Two key eye-tracking metrics—time to first fixation (TTFF) and first fixation duration (FFD)—are harnessed to scrutinize gaze behavior across elements such as wall color, logo signage, wall display fixtures, and media screens. The research unearths statistically significant effects of visual elements on gaze behavior, with particular emphasis on TTFF and FFD. Gender disparities come to light in Cases 2, 3, and 4, affecting FFD on wall color (AOI 1) and TTFF on brand logo signage (AOI 2) in Case 2. Moreover, disparities in design background surface in Cases 1 and 3. Complementing the eye-tracking data and post-experiment interviews capture users' initial gaze attraction and preferences, offering valuable insights into their rationale. In essence, this study underscores the transformative potential of VR technology and eye-tracking techniques in HCI and furnishes actionable insights for those seeking to elevate brand recognition and consumer engagement within immersive virtual retail settings.

Abstract:In this contribution, an analysis of the effect of the adoption of virtual reality on human attention is presented. Specifically, we analyzed whether the use of virtual reality leads to a higher level of attention with respect to the use of the same application on a 2D display system. For this purpose, a subjective experiment based on the Stroop test has been implemented. The analysis performed on the collected data suggests that the immersive virtual reality experience helps the user to focus, thus increasing user performance and reducing the impact of external distractions. The heart rate of the observers was also measured during the experiment. Tests show that the heart rate tends to be higher and more regular when using a virtual reality headset than when using a 2D screen. This may indicate greater user engagement.
