Abstract:It is significant to predict the remaining useful life (RUL) of the bearing to ensure its safe and stable operation. At present, the data-driven method has been successfully applied in the field of bearing RUL prediction. However, the feature correlations between data at different moments may be different, few methods can dynamically identify the change of the feature correlations between input data at different moments, which can impact the performance of the prediction. This article proposes an innovative RUL prediction method based on the adaptive feature correlations aggregation module (AFCA) and gated recurrent unit (GRU) to address this issue. First, statistical features are extracted from the vibration signal, and the fully connected graph is constructed to map the vibration signal data into the graph structure. Subsequently, the AFCA module is designed and constructed, and the AFCA-GRU model is built by combining GRU. A series of constructed fully connected graphs are fed into the model, and the hidden degradation information in graph structure data is mined to realize the prediction of bearing RUL. Among them, AFCA is used to adaptively explore the spatial correlations between graph node features at different moments, and GRU is used to explore the temporal correlations between graph structures. The PHM2012 Challenge dataset is utilized to validate the effectiveness of the proposed method. The comparative experimental results demonstrate that the performance of the method proposed herein surpasses that of other data-driven methodologies, with the capability to accurately predict the RUL of bearings.

Abstract:Effective remaining useful life (RUL) prediction of bearings is essential for the predictive maintenance of rotating machinery. However, the effectiveness of many existing RUL prediction methods depends on expert experience and signal processing algorithms, which limiting the application of these methods in real-life scenarios. This study proposes a novel end-to-end deep learning framework consisting of a multi-scale attention-based dilated causal convolutional (MADCC) module and a multi-layer temporal convolutional network (MTCN) to predict the RUL of bearings using raw vibration data. First, the MADCC module extracts multi-scale temporal features of the bearing degradation process (BDP) and provides fused feature vectors containing comprehensive BDP information for the MTCN module. Subsequently, the MTCN module mines deep temporal dependencies hidden in the fused feature vector to predict the RUL of bearings. Ablation experiments are conducted to analyze the contribution of the framework's components. Three evaluation metrics (root mean square error (RMSE), mean absolute error (MAE), and coefficient of determination (R2)) are used to verify the effectiveness of the proposed framework and other state-of-the-art methods on two public bearing datasets. The experimental results show that the proposed framework achieves the lowest RMSE and MAE and the highest R2, demonstrating excellent performance and potential for RUL prediction of bearings.

Abstract:s: As a pivotal element within the drive system of mechanical equipment, the Remaining Useful Life (RUL) of rolling bearings not only dictates the lifespan of the equipment's drive system but also the overall machine. An inaccurate prediction of the RUL of rolling bearings could hinder the formulation of maintenance strategies and lead to a chain of failures stemming from bearing malfunction, culminating in potentially catastrophic accidents. This paper designs a novel Temporal Convolutional Network-Multi-head Self-Attention (TCN-MSA) model for predicting the RUL of rolling bearings. This model considers the intricate non-linearity and complexity of mechanical equipment systems. It captures long-term dependencies using the causally inflated convolutional structure within the Temporal Convolutional Network (TCN) and simultaneously extracts features from the frequency domain signal. Subsequently, by employing the Multi-head Self-Attention (MSA) mechanism, the model discerns the significance of different features throughout the degradation process of rolling bearings by analyzing global information. The final prediction for rolling bearings' RUL has been successfully attained. To underline the excellence of the method presented in this paper, a comparative analysis was performed with existing methods, such as Convolutional Neural Network (CNN), Gate Recurrent Unit (GRU), and Temporal Convolutional Network (TCN). The results highlight that the model designed in this paper surpasses other existing methods in predicting the RUL of rolling bearings, demonstrating superior prediction accuracy and robust generalization capability.

Abstract:The accurate prediction of the remaining useful life (RUL) of rolling bearings is of immense importance in ensuring the safe and smooth operation of machinery and equipment. Although the prediction accuracy has been improved by a predictive model based on deep learning, it is still limited in engineering because lots of models use single-scale features to predict and assume that the degradation data of each bearing has a consistent distribution. In this paper, A deep convolutional migration network based on spatial pyramid pooling (SPP-CNNTL) is proposed to obtain higher prediction accuracy with self-extraction of multi-feature from the original vibrating signal. And to consider the differences of the data distribution in different failure types, transfer learning (TL) added with maximum mean difference (MMD) measurement function is used in the RUL prediction part. Finally, the data of IEEE PHM 2012 Challenge is used for verification, and the results show that the method in this paper has high prediction accuracy.

Abstract:Deep-learning (DL)-based remaining useful life (RUL) prognostics have achieved prominent advancements to maintain the reliability and safety of industrial equipment. The run-to-failure condition monitoring data of machinery generally takes the form of a long life-cycle sequence containing long and short-term latent degradation patterns, which requires DL models possessing both global and local modeling abilities for RUL prediction. Nevertheless, most existing DL approaches are still inadequate for capturing precise long-time dependencies and grasping local information synchronously. To address this challenge, this article proposes a novel multiscale temporal convolutional transformer (MTCT) to simultaneously extract long-term degradation features and local contextual associations directly from raw monitoring data. It has two distinctive characteristics. First, a convolutional self-attention (CsA) mechanism is developed to insert dilated causal convolution (DCC) into the self-attention mechanism so that the modeling of local context can be incorporated into global modeling to capture more accurate long-term dependency coupling and mitigate the influences of stochastic noises. Second, a temporal convolutional network (TCN) attention module combing TCN and squeeze-and-excitation (SE) attention is designed to select more important degradation-relation features and improve the local representation learning ability. Afterward, an end-to-end RUL prognostic framework based on the MTCT is established for bearings. Comparative studies and ablation experiments are carried out on a real-world dataset of bearings to demonstrate the effectiveness and superiority of the proposed method.

Abstract:In response to the problems of difficult identification of degradation stage start points and inadequate extraction of degradation features in the current rolling bearing remaining life prediction method, a rolling bearing remaining life prediction method based on multi-scale feature extraction and attention mechanism is proposed. Firstly, this paper takes the normalized bearing vibration signal as input and adopts a quadratic function as the RUL prediction label, avoiding identifying the degradation stage start point. Secondly, the spatial and temporal features of the bearing vibration signal are extracted using the dilated convolutional neural network and LSTM network, respectively, and the channel attention mechanism is used to assign weights to each degradation feature to effectively use multi-scale information. Finally, the mapping of bearing degradation features to remaining life labels is achieved through a fully connected layer for the RUL prediction of bearings. The proposed method is validated using the PHM 2012 Challenge bearing dataset, and the experimental results show that the predictive performance of the proposed method is superior to that of other RUL prediction methods.

Abstract:Data-driven machine learning for rolling bearing remaining useful life (RUL) prediction is a promising method in condition-based maintenance. However, due to the uncertainty of optimal hyperparameter tuning of the machine learning model, it is very difficult for a data-driven method to accurately predict the remaining useful life of rolling bearings. Aiming to address this problem, this paper proposes a hybrid model-based on continuous wavelet transform (CWT), convolutional neural network (CNN), Bayesian network (BN) and long short-term memory network (LSTM) for estimating the remaining usage of rolling bearings lifetime. Firstly, the one-dimensional vibration signal of a bearing is divided into six segments and then it is converted into the corresponding two-dimensional time-frequency feature images via CWT. Secondly, the two-dimensional images are input into the two-dimensional CNN for deep feature extraction in order to obtain a series of one-dimensional feature vectors. Finally, it is input into a Bayesian-optimized long short-term memory (BayesianLSTM) model to obtain a prediction of the remaining useful life of the bearing. The effectiveness of the proposed method is verified using bearing data. The verification results show that the proposed method has better prediction accuracy than the other two compared prediction methods, which indicates that the proposed method can effectively extract the bearing fault features and accurately predict the remaining useful life of rolling bearings.

Abstract:The vibration signal characteristics of rolling bearings are closely related to the performance decay process, predicting the remaining useful life (RUL) of rolling bearings by vibration signals can effectively prevent the occurrence of bearing failures. In this paper, a deep learning-based method for rolling bearing RUL prediction is proposed. The convolutional neural network (CNN), which is more effective in extracting local information, is combined with the Transformer structure, which is specialized in extracting global information, to deeply explore the complex mapping relationship between signal features in wavelet power spectrogram and bearing RUL. Meanwhile, the method of detecting the first prediction time of rolling bearings based on 3 σ criteria is improved. The proposed method is validated with the XJTU-SY rolling element bearing accelerated life test datasets, as well as compared with other methods to prove its superiority. The results show that the proposed method can effectively extract bearing degradation information and realize the accurate prediction of rolling bearing RUL. The performance-improved rolling bearing RUL prediction model is highly robust and generalizable, which applies to other mechanical parts performance prediction and can be realized for practical applications in industrial fields.

Abstract:The rolling bearing prognostics holds a great potential in improving maintenance actions and promoting reliability for the operation of the machinery. This paper proposes a novel direct bearing remaining useful life (RUL) prediction approach based on the newly developed temporal convolutional networks (TCN). Unlike many exist data-driven approaches which apply complex feature engineering to achieve efficient results, such as time-frequency analysis and feature selection,etc., the proposed end-to-end prediction approach focus on performing the feature learning more directly and lightly from the raw vibration signals. For the first, signal segmentation is conducted and some statistical features can be attained. Then, these features are fed into the TCN model for RUL prediction. Numerical experiments based on practical rolling bearing dataset show that the proposed approach can not only achieve competitive prediction accuracy, but also require much less time for training in comparison with several baseline data-driven approaches.

Abstract:In industrial applications, nearly half the failures of motors are caused by the degradation of rolling element bearings (REBs). Therefore, accurately estimating the remaining useful life (RUL) for REBs is of crucial importance to ensure the reliability and safety of mechanical systems. To tackle this challenge, model-based approaches are limited by the complexity of mathematical modeling. Conventional data-driven approaches, on the other hand, require massive efforts to extract the degradation features and construct the health index. In this article, a novel data-driven framework is proposed to exploit the adoption of deep convolutional neural networks (CNNs) in predicting the RULs of bearings. More concretely, raw vibrations of training bearings are first processed using the HilbertHuang transform to construct a novel nonlinear degradation energy indicator which can be used as the training label. The CNN is then employed to identify the hidden pattern between the extracted degradation energy indicator and the raw vibrations of training bearings, which makes it possible to estimate the degradation of the test bearings automatically. Finally, testing bearings RULs are predicted through using an $\epsilon$-support vector regression model. The superior performance of the proposed RUL estimation framework, compared with the state-of-the-art approaches, is demonstrated through the experimental results. The generality of the proposed CNN model is also validated by performance test on other bearings undergoing different operating conditions.

Abstract:As the fundamental component of a motor, bearings primarily serve the roles of supporting the guide shaft, minimizing equipment friction, and facilitating interconnections among various equipment. The accurate prediction of bearings’ remaining useful life (RUL) assumes paramount significance in the broader domains of system status maintenance and health management. Presently, deep learning models exhibit automatic feature acquisition capabilities and deliver commendable results in predicting RUL. However, these models tend to overlook the slow-changing dynamics of low-frequency information embedded within mechanical dynamic behavior. To address the aforementioned challenges, we propose a novel approach: an RUL prediction model that incorporates slow feature analysis-assisted attention mechanism with dual long short-term memory (dual-LSTM) networks. This approach enables the simultaneous extraction of slow-changing dynamics and temporal dynamics from measurements, resulting in a more accurate RUL estimation. First, slow-changing features are decomposed on the basis of the automatic features extracted by the autoencoding model, enhancing the ability to capture the overall trend of changes in the full-life cycle of the rolling bearing. Second, an attention mechanism is introduced into the dual-LSTM network, amplifying the significance of key input features while attenuating the influence of irrelevant attributes. The maximum mean discrepancy loss is incorporated into the loss function to mitigate the distribution differences between the training and test datasets. The effectiveness and superiority of the algorithm are validated using the IEEE 2012 PHM challenge and ALT-1A datasets. The results indicate that the proposed approach can offer a slow-changing dynamics perspective on the degradation process of bearings and outperforms existing methods, providing a novel solution for RUL prediction.

Abstract:In the context of predicting the remaining useful life (RUL) of rolling bearings, many models often encounter challenges in identifying the starting point of the degradation stage, and the accuracy of predictions is not high. Accordingly, this paper proposes a technique that utilizes particle swarm optimization (PSO) in combination with the fusing of a one-dimensional convolutional neural network (CNN) and a multihead self-attention (MHSA) bidirectional long short-term memory (BiLSTM) network called PSO-CNN-BiLSTM-MHSA. Initially, the original signals undergo correlation signal processing to calculate the features, such as standard deviation, variance, and kurtosis, to help identify the beginning location of the rolling bearing degradation stage. A new dataset is constructed with similar degradation trend features. Subsequently, the particle swarm optimization (PSO) algorithm is employed to find the optimal values of important hyperparameters in the model. Then, a convolutional neural network (CNN) is utilized to extract the deterioration features of rolling bearings in order to predict their remaining lifespan. The degradation features are inputted into the BiLSTM-MHSA network to facilitate the learning process and estimate the remaining lifespan of rolling bearings. Finally, the degradation features are converted to the remaining usable life (RUL) via the fully connected layer. The XJTU-SY rolling bearing accelerated life experimental dataset was used to verify the effectiveness of the proposed method by k-fold cross-validation. After comparing our model to the CNN-LSTM network model and other models, we found that our model can achieve reductions in mean absolute error (MAE), root mean square error (RMSE), and mean absolute percentage error (MAPE) of 9.27%, 6.76%, and 2.35%, respectively. Therefore, the experimental results demonstrate the model's accuracy in forecasting remaining lifetime and support its ability to forecast breakdowns.

Abstract:Accurate prediction of the remaining useful life (RUL) of rolling bearings is important to ensure the safe operation of mechanical system and to formulate maintenance strategies. Accordingly, this paper proposes a RUL prediction method combining a dilated causal convolutional DenseNet (DCCDenseNet) and an exponential model, and the keys to its implementation include the construction of health indicators that can characterize performance degradation and the determination of first prediction time (FPT). First, continuous wavelet transform is applied to transform time-domain signals into time-frequency images as the input of the network model. Second, a DCCDenseNet model is constructed by introducing the dilated causal convolution into a DenseNet model, which is used to construct health indicators from time-frequency images. It not only inherits the advantages of the DenseNet model, but can also capture the temporal patterns of time series. Finally, an indicator is constructed by using four time-domain statistical indicators to determine the FPT, and it is combined with an exponential model to fit the obtained health indicators to predict RUL. Two rolling bearing datasets are applied to analyze the availability of the suggested method, and its good performance in the RUL prediction is demonstrated by comparing with the results of other methods.

Abstract:Remaining useful life (RUL) prediction is of great importance to improve the reliability and availability of machinery. Traditional rolling bearing RUL prediction methods ignore the impact of bearing degradation states recognition on accurate the RUL prediction. A novel deep learning-based two-stage RUL prognostic approach is presented in this paper by using fast search and find of density peaks clustering (FSFDPC) and multi-dimensional deep neural network (MDDNN). In the first stage, health states of the rolling bearing are automatically perceived by the FSFDPC, where no manual parameters need to be preset. In the second stage, MDDNN is constructed with parallel BLSTM and BGRU channels to extract the multi-dimensional feature maps from the input for accurate RUL prediction. The effectiveness of the proposed two-stage prognostic approach is validated by rolling bearing experimental data of three cases. The comparisons with other existing approaches show that the proposed approach has superior prediction performance under different working conditions.

Abstract:Maintaining the reliability of rotating machinery in industrial environments entails significant challenges. The objective of this paper is to develop a methodology that can accurately predict the condition of rotating machinery in order to facilitate the implementation of effective preventive maintenance strategies. This article proposed a novel RUL-centric data augmentation method, designated as DF-MDAGRU, for the purpose of predicting the remaining useful life (RUL) of bearings. This model is based on an encoder–decoder framework that integrates time–frequency domain feature enhancement with multidimensional dynamic attention gated recurrent units for feature extraction. This method enhances time–frequency domain features through the Discrete Wavelet Downsampling module (DWD) and Convolutional Fourier Residual Block (CFRB). This method employs a Multiscale Channel Attention Module (MS-CAM) and a Multiscale Convolutional Spatial Attention Mechanism (MSSAM) to extract channel and spatial feature information. Finally, the output predictions are processed through linear regression to achieve the final RUL estimation. Experimental results demonstrate that the proposed method outperforms other state-of-the-art approaches on the FEMETO-ST and XJTU datasets.

Abstract:Deep learning has achieved numerous breakthroughs in bearing predicting remaining useful life (RUL). However, the current mainstream deep learning framework inevitably has flaws, including the disadvantage of the small receptive field, the difficulty of learning long-term dependencies and the singularity of feature extraction domains, etc. Given the challenges mentioned above, we propose a new convolutional dual-channel Transformer network (CDCT) for remaining useful life prediction of rolling bearings. In the CDCT, the causal convolution operation is applied to extract local features from the time and frequency domains and add positional encoding to the input signal, while the transformer block is utilized for extracting bidirectional features and fusing them. The CDCT not only has a global receptive field but also can learn long-term dependencies regardless of sequence length. Besides, the time window concatenation is adopted to ameliorate the problem of large amounts of trainable parameters of the Transformer-based models. In the experiments, we conduct a detailed analysis of each crucial element and hyperparameter of the CDCT and compare it to multiple basic and advanced methods. The experimental results highlight the superiority of the CDCT in bearing RUL prediction and demonstrate the effectiveness of crucial elements in the CDCT.

Abstract:Purpose This study aims to introduce a method for predicting the remaining useful life (RUL) of bearings based on parallel feature extraction. The proposed model provides prior knowledge and removes redundant handcrafted feature information, additionally, which focuses on the important features at different time scales. Design/methodology/approach Distinct from traditional parallel feature extraction methods, which can lead to information redundancy, a one-dimensional convolutional autoencoder is introduced to process selected indicators to remove redundancy and retain useful feature information. To fully capture the important degradation information within different stages in the feature sequences, a novel multi-scale attention feature fusion module is proposed to extract degradation features at different time scales. Considering the impact of degradation modes on RUL prediction, a dual-task prediction module based on no degradation mode labels is designed to obtain accurate RUL. Findings Comparative experiments and ablation studies on the PHM2012 bearing dataset verified the effectiveness of the proposed method. Furthermore, the rationality of the selected parameters is confirmed through model parameter analysis. Originality/value The novelty of the proposed method is that it not only provides prior knowledge but also further removes redundant information from prior knowledge. In addition, the distribution differences between the original features and their multi-scale convolution results are measured through Kullback–Leibler divergence as the attention scores, which allows the proposed method to focus on important information at different time scales.
A Novel Combination Neural Network Based on ConvLSTM-Transformer for Bearing Remaining Useful Life Prediction

Abstract:A sensible maintenance strategy must take into account the remaining usable life (RUL) estimation to maximize equipment utilization and avoid costly unexpected breakdowns. In view of some inherent drawbacks of traditional CNN and LSTM-based RUL prognostics models, a novel combination model of the ConvLSTM and the Transformer, which is based on the idea of "Extracting spatiotemporal features and applying them to RUL prediction", is proposed for RUL prediction. The ConvLSTM network can directly extract low-dimensional spatiotemporal features from long-time degradation signals. The Transformer, based entirely on attention mechanisms, can deeply explore the mapping law between deep-level nonlinear spatiotemporal feature information and equipment service performance degradation. The proposed approach is validated with the whole-life degradation dataset of bearings from the PHM 2012 Challenge dataset and the XJTU-SY public dataset. The detailed comparative analysis shows that the proposed method has higher RUL prediction accuracy and outstanding comprehensive prediction performance.

Abstract:Due to the complex and diverse operating conditions of rolling bearings, it is difficult to accurately predict remaining useful life (RUL) of rolling bearings via traditional prediction models. Besides, when a rolling bearing malfunctions, only single channel or single-domain degradation information is considered to bear RUL prediction, and the prediction effect of existing RUL prediction methods is greatly limited. Therefore, in order to address the above issue, a novel method abbreviated as CNN-GRU-MSA with multi-channel feature fusion is proposed for RUL prediction of rolling bearings. Firstly, the statistical features related to the time series are calculated, and the similarity features are constructed based on the obtained statistical features. Then, the sensitive features are selected and fused through specific indicators. Finally, the dual-channel feature fusion is performed to construct a health indicator (HI), which is input into the proposed CNN-GRU-MSA model for training and achieving RUL prediction of rolling bearings. The effectiveness of the proposed method is validated using two benchmark datasets (i.e. IEEE PHM 2012 challenge datasets and XJTU-SY datasets). Experimental results demonstrate the superiority and effectiveness of the proposed method over other similar prediction methods in bearing RUL prediction.

Abstract:The performance of bearings plays a pivotal role in determining the dependability and security of rotating machinery. In intricate systems demanding exceptional reliability and safety, the ability to accurately forecast fault occurrences during operation holds profound significance. Such predictions serve as invaluable guides for crafting well-considered reliability strategies and executing maintenance practices aimed at enhancing reliability. In the real operational life of bearings, fault information often gets submerged within the noise. Furthermore, employing Long Short-Term Memory (LSTM) neural networks for time series prediction necessitates the configuration of appropriate parameters. Manual parameter selection is often a time-consuming process and demands substantial prior knowledge. In order to ensure the reliability of bearing operation, this article investigates the application of three advanced techniques—Maximum Correlation Kurtosis Deconvolution (MCKD), Multi-Scale Permutation Entropy (MPE), and Long Short-Term Memory (LSTM) recurrent neural networks—for the prediction of the remaining useful life (RUL) of rolling bearings. The improved sparrow search algorithm (ISSA) is employed for configuring parameters in the Long Short-Term Memory (LSTM) network. Each technique’s principles, methodologies, and applications are comprehensively reviewed, offering insights into their respective strengths and limitations. Case studies and experimental evaluations are presented to assess their performance in RUL prediction. Findings reveal that MCKD enhances fault signatures, MPE captures complexity, and LSTM excels in modeling temporal patterns. The root mean square error of the prediction results is 0.007. The fusion of these techniques offers a comprehensive approach to RUL prediction, leveraging their unique attributes for more accurate and reliable predictions.
