Abstract:Contamination of aflatoxins has important effect on the quality of corn seed. In this study, hyperspectral imaging technology was used to detect aflatoxin B1 (AFB1) with different concentrations (100, 50, 30, 20 and 10 μg/kg) on corn seeds. The near-infrared hyperspectral data, which were collected from the corn seed samples, were processed by image segmentation method. Then, the spectra in the range of 460–929 nm in the region of seed embryo were extracted from the seed-embryo hyperspectral image. Next, the modeling performance of two schemes under four preprocessing methods (none, multiplicative scatter correction (MSC), standard normal variate (SNV), and 5–3 smoothing), four feature wavelength extraction methods (full wavelength, principal component analysis (PCA), X-loading, and successive projection algorithm (SPA)) and three chemometrics methods (k-nearest neighbor (KNN), linear discriminant analysis (LDA), and support vector machine (SVM)) were compared. The optimal result of the testing set is in the case of “5–3 smoothing” pretreatment, SPA method, and SVM model, with 84.1%, 77.8% and 87.3%, 83.0% accuracies of the training set and testing set respectively in scheme 1 and scheme 2. The optimal accuracy of the testing set obtained by “SPA method” is 3.5% higher than in the case of “full wavelength” method, reducing the model calculations and improving the model accuracy to a certain extent. These 10 wavelengths (460.41, 491.50, 594.72, 617.60, 679.77, 726.69, 739.00, 772.43, 926.10, and 929.03 nm) obtained by “SPA method” provide the possibility for real-time online monitoring AFB1 contamination on corn seeds in the future.
Quantitative aflatoxin B1 detection and mining key wavelengths based on deep learning and hyperspectral imaging in subpixel level

Abstract:Aflatoxin is a serious threat to agricultural safety and human health. This study used a one-dimensional convolutional network to detect peanut aflatoxin B1 content and mine the aflatoxin key wavelengths based on spectral information. First, predicting AFB1 content performance was compared between single-branch and dual-branch convolutional networks. Pearson correlation coefficient of the dual-branch network was 0.77 for toxin content prediction, which was better than the single-branch network model. Then, the key wavelengths of deep learning mining were evaluated using support vector machines under different training folds. The experimental results showed that the key wavelength was optimal with 8 training folds. Finally, deep learning and traditional methods were performed to mine the key wavelengths. The experimental results indicated that the key wavelengths mined by deep learning were better than the traditional method, and the accuracy of deep learning was 91.30% in the test set. The most important wavelength of deep learning was 445 nm. The study indicated that the model accurately predicted toxin content and selected key wavelengths. The model provides an effective method for aflatoxin rapid detection.

Abstract:The oxygen-atom-transfer (OAT) from [(t)BuOCO]Cr(V)(O)(THF) (2) (where (t)BuOCO = [2,6-C(6)H(3)(6-(t)BuC(6)H(3)O)(2)](3-), THF = tetrahydrofuran) to triphenylphosphine (PPh(3)) in THF produces [(t)BuOCO]Cr(III)(THF)(3) (1) and triphenylphosphine oxide (OPPh(3)) at a rate of 69.5(±1.9) M(-1) s(-1) (22 °C). Identical rate constants were attained when acetonitrile (MeCN) and dichloromethane/THF (CH(2)Cl(2)/THF) were used as solvents. Electron paramagnetic resonance (EPR) data shows that the six-coordinate complex, [(t)BuOCO]Cr(V)(O)(THF)(2) (2a) forms upon addition of THF to 2, suggesting 2a as the active OAT species in THF. Similarly, addition of OPPh(3) has no influence on the rate of OAT, but the addition of triphenylphosphorus ylide (CH(2)PPh(3)) to form [(t)BuOCO]Cr(V)(O)(CH(2)PPh(3)) (4) prevents OAT to PPh(3). In CH(2)Cl(2), a [Cr(IV)](2)(μ-O) intermediate forms during the OAT from 2 to PPh(3). The OAT from {[(t)BuOCO]Cr(IV)(THF)}(2)(μ-O) (3) to PPh(3) reveals a zero-order dependence in PPh(3) indicating the dimer must first dissociate prior to OAT. The decay of 3versus time does not follow first-order kinetics due to the formation of a [(t)BuOCO]Cr(III)(THF) species (5) that inhibits the dissociation of 3. The change in concentration of 3versus time during OAT was simulated to obtain approximate rate constants.
A Preliminary Study of Aflatoxin B1 Detection in Peanut Oil by Terahertz Time-Domain Spectroscopy

Abstract:Aflatoxins are fungal secondary toxic metabolites that can cause serious health problems in animals and humans. Terahertz (THz) spectroscopy is promising as a nondestructive analytical tool for chemical and biochemical detection. In this technical note, THz time-domain spectroscopy (THz-TDS) was used for the quantitative analysis of aflatoxin B1 (AFB1) in peanut oil. Chemometrics methods including partial least squares regression (PLSR) and stepwise multiple linear regression (SMLR) were used to build quantitative models. Their performance was compared using two spectral pretreatment methods (first and second derivative). The results show that the SMLR model was more stable than the PLSR model, although its prediction precision was slightly lower. When 1.11 and 0.72 THz frequencies were used, the root mean square errors of calibration (RMSEC) and cross-validation (RMSECV) were 18.2 and 27.7 ppm, respectively, and the corresponding correlation coefficients (r(c) and r(cv)) were 0.9639 and 0.9309, respectively. The overall results indicate that THz-TDS combined with frequency selection could be applied as a rapid and nondestructive tool for the determination of AFB1 content in peanut oil.

Abstract:The visible/near-infrared (Vis/NIR) spectroscopy technique has been widely used for the online detection of soluble solids content (SSC) in apples. However, external factors such as sample size and detection position can cause spectral distortion, resulting in a decline in detection accuracy. In this study, we aimed to develop a more robust prediction model that can resist the impact of sample size and detection position on the model. Firstly, we collected and analyzed the transmission spectra of apple samples under different sizes and detection positions using a self-designed Vis/NIR spectroscopy online acquisition device. It was found that the effect of fruit size and detection position on Vis/NIR spectra was due to optical path difference. Thus, a diameter correction method was utilized to uniformly correct the obtained absorbance spectra. The performance of local models achieved better results after correction. And then, global models with various preprocessing methods were developed. To further improve the model performance, changeable size moving window (CSMW) and competitive adaptive reweighted sampling (CARS) were utilized to select the effective wavelengths. After that, one dimensional-convolutional neural network (1D-CNN) model was constructed, which outperformed the other models without any preprocessing and optimization methods, and the values of RCal2, RMSEC, RPre2, and RMSEP are 0.953, 0.254 %, 0.900, and 0.371 %, respectively. In this study, conventional PLSR modelling methods and deep 1D-CNN method were compared under the influence of the two external factors, and the result showed that 1D-CNN can serve as a more convenient alternative for apple online SSC determination, which could significantly reduce the complexity of the Vis/NIR spectroscopy modeling process.

Abstract:Cotton diseases cause low cotton production and fiber quality. Disease detection methods based on deep learning can integrate feature extraction and improve identification accuracy. We present an automatic cotton disease detection method to improve the identification accuracy of cotton disease. Cotton images are collected using a quadruped robot. ConvNeXt integrates the convolution neural network architecture with intrinsic superiority of transformer. The multiscale spatial pyramid attention (MSPA) module can help ConvNeXt concentrate on important regions of feature maps. ConvNeXt with the MSPA module shows the best recognition results of 97.2%, 99.7% and 100.0% on one competition dataset and two cotton datasets, respectively, with little increase in inference time. It indicates that the proposed model performs well in recognition accuracy with fast detection speed.

Abstract:This work provides a novel approach to monitor the aflatoxin B1 (AFB1) content in maize by near-infrared (NIR) spectra-based deep learning models that integrates Markov transition field (MTF) image coding and a convolutional neural network (CNN) strategy. According to the data structure characteristics of near-infrared spectra, new structures of one-dimensional CNN (1D-CNN) and two-dimensional MTF-CNN (2D-MTF-CNN) were designed to construct a deep learning model for the monitoring of AFB1 in maize. The results obtained showed that compared with the 1D-CNN model, the performance of the 2D-MTF-CNN model had been significantly improved, and its root mean square error of prediction, coefficient of predictive determination, and relative percent deviation were 1.3591 μg·kg−1, 0.9955, and 14.9386, respectively. The results indicate that the MTF is an effective data encoding technique for converting one-dimensional spectra into two-dimensional images. It more intuitively reflects the intrinsic characteristics of the NIR spectra from a new perspective and provides richer spectral information for the construction of deep learning models, which can ensure the detection accuracy and generalization performance of deep learning quantitative detection models. This study provides a new analytical perspective for the chemometrics analysis of the NIR spectroscopy.

Enhanced detection of Aspergillus flavus in peanut kernels using a multi-scale attention transformer (MSAT): Advancements in food safety and contamination analysis

Abstract:In this study, a multi-scale attention transformer (MSAT) was coupled with hyperspectral imaging for classifying peanut kernels contaminated with diverse Aspergillus flavus fungi. The results underscored that the MSAT significantly outperformed classic deep learning models, due to its sophisticated multi-scale attention mechanism which enhanced its classification capabilities. The multi-scale attention mechanism was utilized by employing several multi-head attention layers to focus on both fine-scale and broad-scale features. It also integrated a series of scale processing layers to capture features at different resolutions and incorporated a self-attention mechanism to integrate information across different levels. The MSAT model achieved outstanding performance in different classification tasks, particularly in distinguishing healthy peanut kernels from those contaminated with aflatoxigenic fungi, with test accuracy achieving 98.42±0.22%. However, it faced challenges in differentiating peanut kernels contaminated with aflatoxigenic fungi from those with non-aflatoxigenic contamination. Visualization of attention weights explicitly revealed that the MSAT model's multi-scale attention mechanism progressively refined its focus from broad spatial-spectral features to more specialized signatures. Overall, the MSAT model's advanced processing capabilities marked a notable advancement in the field of food quality safety, offering a robust and reliable tool for the rapid and accurate detection of Aspergillus flavus contaminations in food.

Abstract:In this study, a novel uniform manifold approximation and projection combined-improved simultaneous optimization genetic algorithm-convolutional neural network (UMAP-ISOGA-CNN) algorithm was proposed. The improved simultaneous optimization genetic algorithm (ISOGA) combined with convolutional neural network (CNN) to optimize the architecture, hyperparameters, and optimizer of the CNN model simultaneously. Additionally, a uniform manifold approximation and projection (UMAP) method was used to visualize the feature space of all feature layers of the ISOGA-CNN model. The UMAP-ISOGA-CNN algorithm combined with visible and near-infrared hyperspectral imaging was used to identify peanut kernels contaminated with Aspergillus flavus and to distinguish their storage time, which is essential for the food industry to monitor the freshness of products. Overall, the UMAP-ISOGA-CNN algorithm provides useful insights into the feature space of the ISOGA-CNN model, contributing to a better understanding of the model's internal mechanisms. This study has practical implications for the food industry and future research on deep learning optimization.

Abstract:This study designs a chemometric framework for quantitatively evaluating aflatoxin B 1 (AFB 1 ) in peanuts based on near-infrared (NIR) spectroscopy technique. The NIR spectra of peanut samples exhibiting diverse fungal contamination levels were acquired using a portable NIR spectrometer. Subsequently, appropriate pre-processing techniques were employed for data refinement. To streamline the analysis, the iterative variable subset optimization (IVSO) technique was employed to conduct an initial screening of the pre-processed NIR spectra, eliminating numerous irrelevant variables. Building upon this screening process, the beluga whale optimization (BWO) algorithm was utilized to optimize the selected feature variables further. Subsequently, support vector machine (SVM) models were developed using the refined near-infrared spectral features to test AFB 1 in peanuts quantitatively. The results indicate that the SVM model significantly improves detection performance and generalization proficiency, particularly after secondary optimization using BWO-IVSO. Among the different models considered, the SVM model established after BWO-IVSO optimization exhibited the most extraordinary level of generalization, with a root mean square error of prediction of 24.6322 μg∙kg −1 , a correlation coefficient of 0.9761, and a relative percent deviation of 4.6999. Overall, this investigation highlights the effectiveness of the proposed NIR spectroscopy model based on BWO-IVSO-SVM for quantitatively analyzing AFB 1 in peanuts. The study contributes valuable technical and methodological insights that can serve as a reference for rapidly determining mycotoxins in cereal crops.

Abstract:Aflatoxins in moldy peanuts are seriously toxic to humans. These kernels need to be screened in the production process. Hyperspectral imaging techniques can be used to identify moldy peanuts. However, the changes in spectral information and texture information caused by the difference in moisture content in peanuts will affect the identification accuracy. To reduce and eliminate the influence of this factor, a data augmentation method based on interpolation was proposed to improve the generalization ability and robustness of the model. Firstly, the near-infrared hyperspectral images of 5 varieties, 4 classes, and 3 moisture content gradients with 39,119 kernels were collected. Then, the data augmentation method called the difference of spectral mean (DSM) was constructed. K-nearest neighbors (KNN), support vector machines (SVM), and MobileViT-xs models were used to verify the effectiveness of the data augmentation method on data with two gradients and three gradients. The experimental results show that the data augmentation can effectively reduce the influence of the difference in moisture content on the model identification accuracy. The DSM method has the highest accuracy improvement in 5 varieties of peanut datasets. In particular, the accuracy of KNN, SVM, and MobileViT-xs using the data of two gradients was improved by 3.55%, 4.42%, and 5.9%, respectively. Furthermore, this study provides a new method for improving the identification accuracy of moldy peanuts and also provides a reference basis for the screening of related foods such as corn, orange, and mango.

Abstract:This study described the rapid determination of potential aflatoxigenic fungi contamination on peanut kernels based on headspace-gas chromatography-ion mobility spectrometry (HS-GC-IMS) coupled to fluorescence spectroscopy. Data-level and feature-level fusion strategies were introduced to integrate HS-GC-IMS and fluorescence spectra, aiming at improving the performances of identification and prediction models. The application of feature-level data fusion using first 10 PCs coupled with orthogonal partial least squares discriminant analysis (OPLS-DA) offered more accurate characterization (96.7 %) for aflatoxigenic and non-aflatoxigenic fungal infection on peanut samples. Regression models were established for predicting colony counts of peanuts infected with aflatoxigenic fungi based on independent and fused signals by partial least squares regression (PLSR). Feature-level data fusion using first 10 PCs achieved the best performances in colony counts predictions for A. fiavus (R-2 = 0.950) and A. parasiticus (R-2 = 0.971). These results demonstrated that the combination of HS-GC-IMS and fluorescence spectra might offer the feasibility for early detection of potential aflatoxigenic risk in peanuts.
Identification of fungi-contaminated peanuts using hyperspectral imaging technology and joint sparse representation model

Abstract:Peanuts with fungal contamination may contain aflatoxin, a highly carcinogenic substance. We propose the use of hyperspectral imaging to quickly and noninvasively identify fungi-contaminated peanuts. The spectral data and spatial information of hyperspectral images were exploited to improve identification accuracy. In addition, successive projection was adopted to select the bands sensitive to fungal contamination. Furthermore, the joint sparse representation based classification (JSRC), which considers neighboring pixels as belonging to the same class, was adopted, and the support vector machine (SVM) classifier was used for comparison. Experimental results show that JSRC outperforms SVM regarding robustness against random noise and considering pixels at the edge of the peanut kernel. The classification accuracy of JSRC reached 99.2% and 98.8% at pixel scale, at least 98.4% and 96.8% at kernel scale for two peanut varieties, retrieving more accurate and consistent results than SVM. Moreover, fungi-contaminated peanuts were correctly marked in both learning and test images.
Qualitative and quantitative detection of aflatoxins B1 in maize kernels with fluorescence hyperspectral imaging based on the combination method of boosting and stacking

Abstract:The most widespread, toxic, and harmful toxin is aflatoxins B1 (AFB1). The fluorescence hyperspectral imaging (HSI) system was employed for AFB1 detection in this study. This study developed the under sampling stacking (USS) algorithm for imbalanced data. The results indicated that the USS method combined with ANOVA for featured wavelength achieved the best performance with the accuracy of 0.98 for 20 or 50 μg /kg threshold using endosperm side spectra. As for the quantitative analysis, a specified function was used to compress AFB1 content, and the combination of boosting and stacking was used for regression. The support vector regression (SVR)-Boosting, Adaptive Boosting (AdaBoost), and extremely randomized trees (Extra-Trees)-Boosting were used as the base learner, while the K nearest neighbors (KNN) algorithm was used as the meta learner could obtain the best results, with the correlation coefficient of prediction (R<sub>p</sub>) was 0.86. These results provided the basis for developing AFB1 detection and estimation technologies.

Abstract:Moldy peanut seeds are damaged by mold, which seriously affects the germination rate of peanut seeds. At the same time, the quality and variety purity of peanut seeds profoundly affect the final yield of peanuts and the economic benefits of farmers. In this study, hyperspectral imaging technology was used to achieve variety classification and mold detection of peanut seeds. In addition, this paper proposed to use median filtering (MF) to preprocess hyperspectral data, use four variable selection methods to obtain characteristic wavelengths, and ensemble learning models (SEL) as a stable classification model. This paper compared the model performance of SEL and extreme gradient boosting algorithm (XGBoost), light gradient boosting algorithm (LightGBM), and type boosting algorithm (CatBoost). The results showed that the MF-LightGBM-SEL model based on hyperspectral data achieves the best performance. Its prediction accuracy on the data training and data testing reach 98.63% and 98.03%, respectively, and the modeling time was only 0.37s, which proved that the potential of the model to be used in practice. The approach of SEL combined with hyperspectral imaging techniques facilitates the development of a real-time detection system. It could perform fast and non-destructive high-precision classification of peanut seed varieties and moldy peanuts, which was of great significance for improving crop yields.

Abstract:Red ginseng is widely used in food and pharmaceuticals due to its significant nutritional value. However, during the processing and storage of red ginseng, it is susceptible to grow mold and produce mycotoxins, generating security issues. This study proposes a novel approach using hyperspectral imaging technology and a 1D-convolutional neural network-residual-bidirectional-long short-term memory attention mechanism (1DCNN-ResBiLSTM-Attention) for pixel-level mycotoxin recognition in red ginseng. The "Red Ginseng-Mycotoxin" (R-M) dataset is established, and optimal parameters for 1D-CNN, residual bidirectional long short-term memory (ResBiLSTM), and 1DCNN-ResBiLSTM-Attention models are determined. The models achieved testing accuracies of 98.75%, 99.03%, and 99.17%, respectively. To simulate real detection scenarios with potential interfering impurities during the sampling process, a "Red Ginseng-Mycotoxin-Interfering Impurities" (R-M-I) dataset was created. The testing accuracy of the 1DCNN-ResBiLSTM-Attention model reached 96.39%, and it successfully predicted pixel-wise classification for other unknown samples. This study introduces a novel method for real-time mycotoxin monitoring in traditional Chinese medicine, with important implications for the on-site quality control of herbal materials.

Abstract:Carbachol and norepinephrine induce glycogen breakdown in rat submaxillary glands incubated in vitro. These effects are suppressed by specific inhibitors of cholinergic receptors (atropine, a muscarinic blocker) and of adrenergic receptors (propranolol, a beta-blocker and phentolamine, an alpha-blocker). The beta-adrenergic effect seems to be mediated through the adenosine 3':5'-monophosphate system, whereas the alpha-adrenergic and cholinergic effects are dependent of Ca2+ influx into cell. In the two latter systems, it is suggested that a direct activation of phosphorylase b kinase by calcium takes place. These data clearly indicate that glycogenolysis in rat submaxillary glands in vitro can be independently affected by sympathetic and parasympathetic agents via specific receptors.
Peanut Defect Identification Based on Multispectral Image and Deep Learning

Abstract:To achieve the non-destructive detection of peanut defects, a multi-target identification method based on the multispectral system and improved Faster RCNN is proposed in this paper. In terms of the system, the root-mean-square contrast method was employed to select the characteristic wavelengths for defects, such as mildew spots, mechanical damage, and the germ of peanuts. Then, a multispectral light source system based on a symmetric integrating sphere was designed with 2% nonuniformity illumination. In terms of Faster RCNN improvement, a texture-based attention and a feature enhancement module were designed to enhance the performance of its backbone. In the experiments, a peanut-deficient multispectral dataset with 1300 sets was collected to verify the detection performance. The results show that the evaluation metrics of all improved compared with the original network, especially in the VGG16 backbone network, where the mean average precision (mAP) reached 99.97%. In addition, the ablation experiments also verify the effectiveness of the proposed texture module and texture enhancement module in peanut defects detection. In conclusion, texture imaging enhancement and efficient extraction are effective methods to improve the network performance for multi-target peanut defect detection.

Abstract:Aflatioxin B1 (AFB1) has been recognized by the International Agency of Research on Cancer as a group 1 carcinogen in animals and humans. A fast, batch, and real-time control and no chemical pollution method was developed for the discrimination and quantification prediction of AFB1-infected peanuts by applying Fourier transform near-infrared (FT-NIR) coupled with chemometrics. Initially, the near-infrared transmission (NIRT) and diffuse reflection (NIRR) modules were applied to collect spectra of the samples. The principal component analysis (PCA) method was employed to extract the characteristic wavelength, followed by different preprocessing methods (seven methods) to build an effective linear discriminant analysis (LDA) classification and partial least squares (PLS) quantification models. The results showed that, for both the NIRT or NIRR modules, the LDA classification models satisfactorily distinguished peanuts infected with AFB1 or from those not infected, with external validation showing a 100% correct identification rate and a 0% misjudgment rate. In addition, combined with the concentration of AFB1 in peanuts determined by enzyme-linked immunoassay assay, the best partial least squares (PLS) models were established, with a combination of the first derivative and the Norris derivative filter smoothing pretreatment (Rc2 = 0.937 and 0.984, RMSECV = 3.92% and 2.22%, RPD = 3.98 and 7.91 for NIRR and NIRT, respectively). The correlation coefficient between the predicted value and the reference value in the external verification was 0.998 and 0.917, respectively. This study highlights that both spectral acquisition modules meet the requirements of online, rapid, and accurate identification of peanut AFB1 infection in the early stages.

Abstract:Automated detection and identification of vegetable diseases can enhance vegetable quality and increase profits. Images of greenhouse-grown vegetable diseases often feature complex backgrounds, a diverse array of diseases, and subtle symptomatic differences. Previous studies have grappled with accurately pinpointing lesion positions and quantifying infection degrees, resulting in overall low recognition rates. To tackle the challenges posed by insufficient validation datasets and low detection and recognition rates, this study capitalizes on the geographical advantage of Shouguang, renowned as the "Vegetable Town," to establish a self-built vegetable base for data collection and validation experiments. Concentrating on a broad spectrum of fruit and vegetable crops afflicted with various diseases, we conducted on-site collection of greenhouse disease images, compiled a large-scale dataset, and introduced the Space-Time Fusion Attention Network (STFAN). STFAN integrates multi-source information on vegetable disease occurrences, bolstering the model's resilience. Additionally, we proposed the Multilayer Encoder-Decoder Feature Fusion Network (MEDFFN) to counteract feature disappearance in deep convolutional blocks, complemented by the Boundary Structure Loss function to guide the model in acquiring more detailed and accurate boundary information. By devising a detection and recognition model that extracts high-resolution feature representations from multiple sources, precise disease detection and identification were achieved. This study offers technical backing for the holistic prevention and control of vegetable diseases, thereby advancing smart agriculture. Results indicate that, on our self-built VDGE dataset, compared to YOLOv7-tiny, YOLOv8n, and YOLOv9, the proposed model (Multisource Information Fusion Method for Vegetable Disease Detection, MIFV) has improved mAP by 3.43%, 3.02%, and 2.15%, respectively, showcasing significant performance advantages. The MIFV model parameters stand at 39.07 M, with a computational complexity of 108.92 GFLOPS, highlighting outstanding real-time performance and detection accuracy compared to mainstream algorithms. This research suggests that the proposed MIFV model can swiftly and accurately detect and identify vegetable diseases in greenhouse environments at a reduced cost.
