Abstract:This letter proposes a novel deep learning (DL) approach to resolve the electromagnetic inverse scattering (EMIS) problems. The conventional approaches of resolving EMIS problems encounter assorted difficulties, such as high contrast, high computational cost, inevitable intrinsic nonlinearity, and strong ill-posedness. To surmount these difficulties, a novel DL approach is proposed based on a novel complex-valued deep fully convolutional neural network structure. The proposed complex-valued deep learning model for solving EMIS problems composes of an encoder network and its corresponding decoder network, followed by a final pixel-wise regression layer. The complex-valued encoder network extracts feature fragments from received scattered field data, while the role of the complex-valued decoder network is mapping the feature fragments to retrieve the final contrasts (permittivities) of dielectric scatterers. Hence, the proposed deep learning model functions as an "heterogeneous" transformation process, where measured scattering field data is converted into the corresponding contrasts of scatterers. As a consequence, the EMIS problem could be resolved accurately even for extremely high-contrast targets. Numerical benchmarks have illustrated the feasibility and accuracy of our proposed approach. The proposed approach opens a novel path for the deep learning-based real-time quantitative microwave imaging for high-contrast scatterers.

Abstract:Electromagnetic inverse scattering (EMIS) is uniquely positioned among many inversion methods because it enables to image the scene in a contactless, quantitative and super-resolution way. Although many EMIS approaches have been proposed to date, they usually suffer from two important challenges, i.e., time-consuming data acquisition and computationally -prohibitive data post processing, especially for large-scale objects with high and even moderate contrasts. To tackle the challenges, we here propose a framework of intelligent EMIS with the aid of deep learning techniques and information metasurfaces, enabling to the efficient data acquisition and instant data processing in a smart way. Towards this goal, as illustrative examples, we considerably extend the canonical contrast source inversion (CSI) algorithm, a canonical EMIS method by updating the contrast via the generative adversarial network (GAN), an unsupervised deep learning approach, leading to a novel physics-informed unsupervised deep learning method for EMIS, referred to as CSI-GAN in short. Compared with existing deep learning solutions for EMIS, our method relies on the supervision of physical law instead of the labeled training dataset, beating the bottleneck arising from the collection of labeled training datasets. Furthermore, we propose a scheme of adaptive data acquisition with the use of information metasurface in a cost-efficiency way, remarkably reducing the number of measurements and thus speeding up the data acquisition but maintaining the reconstruction's quality. Illustrative examples are provided to demonstrate the performance gain in terms of reconstruction quality, showing the promising potentials for providing the intelligent scheme for the EMIS problems.

Abstract:Electromagnetic inverse scattering problem (ISP) refers to using the measured field data to reconstruct the physical and geometric properties of the scattering target in the detection area. The ISP is inherently nonlinear, ill-conditioned and noise-afflicted. Traditional iterative optimization methods are unstable, time-consuming, inaccurate, and can easily get trapped in local optimums, making it difficult to achieve high-performance real-time imaging. Recently, the diffusion model in deep learning has become a leading solution in the field of image generation, demonstrating exceptional robustness and immunity to noise. In this paper, we use diffusion model and employ 2D panoramic image as a guiding tool for the 3D model reconstruction of electromagnetic scattering to tackle the aforementioned challenges in ISP. It is an innovative attempt to solve the ISP by using the diffusion model, and it has been well verified in the experimental results.
Nonlinear Electromagnetic Inverse Scattering Using DeepNIS

Abstract:Nonlinear electromagnetic (EM) inverse scattering is a quantitative and super-resolution imaging technique, in which the more realistic interactions between the internal structure of scene and EM wavefield has been taken into account the imaging procedure, in contrast to conventional tomography. However, it poses important challenges arising from its intrinsic strong nonlinearity, ill-posedness and expensive computation costs. In this work, we build the connection between the CNN and the unfold iterative solution to nonlinear electromagnetic inverse scattering, and then establish a novel CNN, termed as DeepNIS, for the nonlinear electromagnetic inverse scattering. The DeepNIS is a non-iterative solution to the nonlinear electromagnetic inverse scattering. A central issue to the DeepNIS-based solution is the convolution operation, which can be implemented in parallel. The noniterative and parallelizable natures of the DeepNIS imaging mechanism make it very suitable for dealing with large-scale inverse scattering problems. We showed that the DeepNIS has the overwhelming advantage over conventional inverse scattering methods in terms of the image quality and computational time. Our experimental results demonstrate that the proposed DeepNIS are capable of learning the inverse mapping between the raw intensity image and object directly from the experimental data. The results also suggest that the neural network can “learn” the governing equations of the system, including its forward operator and possible deviations from underlying idealizations and assumptions. Nonetheless, we still remark that one can explore more advanced CNN architectures to get more impressive inverse scattering results. To summarize, the DeepNIS could remarkably break the limitation of the conventional inverse scattering strategies, and can be used for treating the nonlinear electromagnetic inverse scattering with large-scale and high-contrast objects.

Abstract:Reconstructing the exact electromagnetic property of unknown targets from the measured scattered field is challenging due to the intrinsic nonlinearity and ill-posedness. In this article, a new scheme, named the modified contrast scheme (MCS), is proposed to tackle nonlinear inverse scattering problems (ISPs). A local-wave amplifier coefficient is used to form the modified contrast, which is able to alleviate the global nonlinearity in original ISPs without decreasing the accuracy of the problem formulation. Moreover, the modified contrast is more suitable to be the input of the deep learning scheme, due to the unity bound of the modified contrast. The numerical results show that MCS with the modified contrast input performs well in both 2-D and 3-D testing examples in real time after offline training process, even in high-relative-permittivity cases. Compared with the dominant current scheme, a significant improvement is achieved in reconstructing high-contrast scatterers.

Abstract:The electromagnetic-inverse-scattering (EMIS) problem is solved by a novel two-step deep-learning (DL) approach in this article. The newly proposed two-step DL approach not only predicts the multifrequency EM scattered field, but also overcomes the limitation of the conventional methods for solving EMIS problems, such as expensive computational cost, strong ill-conditions, and invalidity on high contrast. In the first step, the complex-valued deep residual convolutional neural network (DRCNN) is utilized to predict multifrequency EM scattered fields only using single-frequency EM scattered field information. Based on a new complex-valued deep convolutional encoder-decoder (DCED) structure, the second step utilizes the obtained multifrequency EM scattered field "images" to realize the reconstruction of the target scatterers. In such a manner, the proposed approach can solve the EMIS problem accurately and efficiently even for inhomogeneous and high-contrast scatterers. The training of the proposed two DL models is based on the simple synthetic dataset. Numerical examples based on various dielectric objects are given to demonstrate the accuracy and performance of the newly proposed approach. The proposed DL-based method opens a new path for handling real-time quantitative microwave imaging.

Abstract:This paper is devoted to solving a full-wave inverse scattering problem (ISP), which is aimed at retrieving permittivities of dielectric scatterers from the knowledge of measured scattering data. ISPs are highly nonlinear due to multiple scattering, and iterative algorithms with regularizations are often used to solve such problems. However, they are associated with heavy computational cost, and consequently, they are often time-consuming. This paper proposes the convolutional neural network (CNN) technique to solve full-wave ISPs. We introduce and compare three training schemes based on U-Net CNN, including direct inversion, backpropagation, and dominant current schemes (DCS). Several representative tests are carried out, including both synthetic and experimental data, to evaluate the performances of the proposed methods. It is demonstrated that the proposed DCS outperforms the other two schemes in terms of accuracy and is able to solve typical ISPs quickly within 1 s. The proposed deep-learning inversion scheme is promising in providing quantitative images in real time.

Abstract:This paper proposes a novel electromagnetic (EM) inversion solver based on a two-step deep learning (DL) framework. The framework consists of the deep convolutional asymmetric encoder-decoder structure (DCAEDS) followed by the deep residual convolutional neural network (DRCNN). In the first step, DCAEDS utilizes EM scattered field data from a single-frequency one-time measurement to coarsely retrieve the initial contrasts (permittivities) of target scatterers. In the second step, DRCNN employs a mixed input scheme, comprising the initially-reconstructed permittivities from the first step and the original EM scattered field data, to significantly improve the retrieved contrasts (permittivities) and refine the reconstruction of targets. Consequently, the proposed EM inversion solver achieves excellent accuracy and efficiency, even for high-contrast targets. The proposed solver is flexible as it is required only for a single-frequency one-time measurement on the EM scattered field. Moreover, the proposed two-step DL-based solver overcomes the limitations of conventional methods, such as high computational costs and ill-posedness. Numerical benchmarks based on various dielectric objects demonstrate the feasibility of the proposed EM inversion solver, highlighting its potential as a candidate for real-time quantitative EM inversion for high-contrast targets.

Abstract:This article studies the full-wave electromagnetic inverse scattering (EMIS) problem that aims to retrieve the permittivities of dielectric scatterers based on the knowledge of measured scattered fields. A physics-induced deep learning (DL) scheme termed contrastive learning-based subspace optimization and semantic segmentation-assisted reconstruction (CLSO-SSR) is proposed to solve this problem. The proposed CLSO-SSR model is novel in aspects: 1) a contrastive learning network to provide an initial estimate of the contrast source so that both the probability of the local optima and the time consumption of the inversion process are greatly reduced and 2) a semantic segmentation network with an attention mechanism to mitigate the nonlinearity caused by the multiple scattering effects. Extensive numerical experiments are carried out to show that the proposed CLSO-SSR scheme can significantly improve upon the permittivity reconstruction performance as opposed to existing alternatives.

Abstract:This article proposes a novel fast electromagnetic (EM) inversion solver for heterogeneous scatterers with high contrast. In order to ensure inversion accuracy, the conventional solvers for the EM inverse scattering (EMIS) problems usually require EM scattered field information originating from multiple incident EM waves, resulting in tedious measurement operation and considerable measurement data for inversion computation. Thus, the conventional solvers are difficult to suit for real-time quantitative EM problems, which require relatively simple measurement operations and small measurement data dimensions. To overcome these challenges, a novel EM inversion solver is proposed based on a conditional deep convolutional generative adversarial network (CDCGAN). The proposed CDCGAN includes the generator with an EM scattering simulator and the corresponding discriminator, both consisting of complex-valued deep convolutional neural networks (DConvNets). The trained CDCGAN can be successfully applied to inhomogeneous and high-contrast scatterers only by employing one single incident EM wave in single-frequency and far-field measurement, which greatly simplifies measurement and reduces the computation complexity for its further inversion computation. Numerical examples have indicated the accuracy and feasibility of the proposed DL-based inversion solver, which acts as the potential candidate for solving real-time quantitative EM problems.

Abstract:In this paper, to bridge the gap between physical knowledge and learning approaches, we propose an induced current learning method (ICLM) by incorporating merits in traditional iterative algorithms into the architecture of convolutional neural network (CNN). The main contributions of the proposed method are threefold. First, to the best of our knowledge, it is the first time that the contrast source is learned to solve full-wave inverse scattering problems (ISPs). Second, inspired by the basis-expansion strategy in the traditional iterative approach for solving ISPs, a combined loss function with multiple labels is defined in a cascaded end-to-end CNN (CEE-CNN) architecture to decrease the nonlinearity of objective function, where no additional computational cost is introduced in generating extra labels. Third, to accelerate the convergence speed and decrease the difficulties of the learning process, the proposed CEE-CNN is designed to focus on learning the minor part of the induced current by introducing several skip connections and to bypass the major part of induced current to the output layers. The proposed method is compared with the state-of-the-art of deep learning scheme and a well-known iterative ISP solver, where numerical and experimental tests are conducted to verify the proposed ICLM.

Abstract:The solution of electromagnetic (EM) inverse scattering problems is hindered by challenges, such as ill-posedness, nonlinearity, and high computational costs. Recently, deep learning was shown to be a promising tool in addressing these challenges. In particular, it is possible to establish a connection between a deep convolutional neural network (CNN) and iterative solution methods of EM inverse scattering. This led to the development of an efficient CNN-based solution to EM inverse problems, termed DeepNIS. It has been shown that DeepNIS can outperform conventional inverse scattering solution methods in terms of both the image quality and computational time. In this letter, we evaluate the DeepNIS performance as a function of the number of layers using structure similarity index measure and mean square error metrics. In addition, we probe the dynamic evolution behavior of DeepNIS by examining its near-isometry property and show that, after a proper training stage, the proposed CNN has near-optimal stability properties.

Abstract:This work proposes a novel deep learning (DL) framework to solve the electromagnetic inverse scattering (EMIS) problems. The proposed framework integrates the complex-valued deep convolutional neural network (DConvNet) into the supervised descent method (SDM) to realize both off-line training and on-line “imaging” prediction for EMIS. The offline training consists of two parts: 1) DConvNet training: the training dataset is created, and the proposed DConvNet is trained to realize the EM forward process and 2) SDM training: the trained DConvNet is integrated into the SDM framework, and the average descent directions between the initial prediction and the true label of SDM iterative schemes are learned based on the same dataset in part 1). In the online step, the contrasts (permittivities) reconstruction of scatterers is realized by the SDM iteration process based on learned descent directions, while its forward process is achieved by the trained complex-valued DConvNet. Ultimately, this framework provides a new perspective to integrate the prior information into the EMIS solving process with the maintained accuracy. Unlike the conventional SDM, the novel proposed framework can significantly shorten the computation and realize the real-time imaging. Various numerical examples and discussions are provided to demonstrate the efficiency and accuracy of the proposed novel framework.
Multi-frequency Neural Born Iterative Method for Solving 2-D Inverse Scattering Problems

Abstract:In this work, we propose a deep learning-based imaging method for addressing the multi-frequency electromagnetic (EM) inverse scattering problem (ISP). By combining deep learning technology with EM physical laws, we have successfully developed a multi-frequency neural Born iterative method (NeuralBIM), guided by the principles of the single-frequency NeuralBIM. This method integrates multitask learning techniques with NeuralBIM's efficient iterative inversion process to construct a robust multi-frequency Born iterative inversion model. During training, the model employs a multitask learning approach guided by homoscedastic uncertainty to adaptively allocate the weights of each frequency's data. Additionally, an unsupervised learning method, constrained by the physical laws of ISP, is used to train the multi-frequency NeuralBIM model, eliminating the need for contrast and total field data. The effectiveness of the multi-frequency NeuralBIM is validated through synthetic and experimental data, demonstrating improvements in accuracy and computational efficiency for solving ISP. Moreover, this method exhibits strong generalization capabilities and noise resistance. The multi-frequency NeuralBIM method explores a novel inversion method for multi-frequency EM data and provides an effective solution for the electromagnetic ISP of multi-frequency data.

Abstract:In this paper, a new deep learning technique is investigated to improve the solution of electromagnetic inverse scattering problems (ISPs). The basic idea of this technique is to introduce the attention mechanism to U-Net. By doing this, the deep learning model can automatically learn to focus on target areas of the measured scattered field matrix. In this way, the proposed technique can offer higher accuracy and faster convergence compared with the traditional deep learning networks. Numerical results validate the efficacy of the proposed technique.

To tackle these difficulties, we, for the first time to our best knowledge, exploit a connection between the deep neural network (DNN) architecture and the iterative method of nonlinear EM inverse scattering. This enables the development of a novel DNN-based methodology for nonlinear EM inverse problems (termed here DeepNIS). The proposed DeepNIS consists of a cascade of multilayer complex-valued residual convolutional neural network modules. We numerically and experimentally demonstrate that the DeepNIS outperforms remarkably conventional nonlinear inverse scattering methods in terms of both the image quality and computational time. We show that DeepNIS can learn a general model approximating the underlying EM inverse scattering system. It is expected that the DeepNIS will serve as powerful tool in treating highly nonlinear EM inverse scattering problems over different frequency bands, which are extremely hard and impractical to solve using conventional inverse scattering methods.

Abstract:In this paper, two new approaches are presented for the solution of electromagnetic inverse scattering problems when amplitude-only data are available. The proposed techniques are based on a customized version, which are the so-called contrast source inversion (CSI) and multiplicative regularized CSI (MRCSI) methods. In the proposed approaches, denoted as the phaseless-data (PD)-CSI and the PD-MRCSI, only the term of the cost functional concerning the mismatch between the measured and estimated field data (i.e., the data equation) has been properly redefined. Moreover, the back-projection algorithm has been modified to provide an initial solution ensuring the rapid convergence of the optimization procedures and avoid the reconstruction of false solutions. A set of representative results concerning numerical as well as experimental tests is reported to show the accuracy of the proposed amplitude-only reconstruction approaches.

Abstract:Without phase information of the measured field data, the phaseless data inverse scattering problems (PD-ISPs) counter more serious nonlinearity and ill-posedness compared with full data ISPs (FD-ISPs). In this article, we propose a learning-based inversion approach in the frame of the U-net convolutional neural network (CNN) to quantitatively image unknown scatterers located in homogeneous background from the amplitude-only measured total field (also denoted PD). Three training schemes with different inputs to the U-net CNN are proposed and compared, i.e., the direct inversion scheme (DIS) with phaseless total field data, retrieval dominant induced currents by the Levenberg–Marquardt (LM) method (PD-DICs), and PD with contrast source inversion (PD-CSI) scheme. We also demonstrate the setup of training data and compare the performance of the three schemes using both numerical and experimental tests. It is found that the proposed PD-CSI and PD-DICs perform better in terms of accuracy, generalization ability, and robustness compared with DIS. PD-CSI has the strongest capability to tackle with PD-ISPs, which outperforms the PD-DICs and DIS.

The scattering behavior of hybrid dielectric and perfect electric conductors (PEC) scatterers is modeled by the T-matrix method. A rough image of the zero-order T-matrix coefficients for unknown scatterers is first reconstructed by the backpropagation (BP) method, which is then refined by an attention-assisted pix2pix generative adversarial network (GAN). The spatial attention mechanism is utilized to enforce the generator network to learn salient features of the unknown scatterers instead of the background. The adversarial training of the generator and the discriminator further enables the reconstructed image to be constrained by high-level features of reference scatterers. Numerical tests on both synthetic and experimental data verify the superior performance of the proposed method for ISP reconstructions with hybrid scatterers. It effectively expands the application scope of learning-based ISP methods to reconstruct scatterers without knowing the BCs of scatterers in advance.
