Abstract:It is crucial for marine researchers and preservationists to routinely evaluate the relative abundance of fish species in their environments and monitor changes in their populations. Different automated computer-based fish sampling systems in underwater videos have been offered instead of arduous hand sampling. However, no ideal solution exists for automated fish identification and species classification. This is mainly because of the challenges involved in filming underwater, such as varying light levels, fish concealment, changing backgrounds, murky water, limited resolution, intricate backgrounds, fish shape distortions, obstruction from other water bodies, and subtle differences among specific fish species. The proposed method uses an improved vision transformer (IMViT) for detection and classification. To capture the inductive bias information from images, the traditional ViT model incorporates the convolutional and residual units of ResNet to improve the architecture of the ViT model when working with a small-scale dataset. Our results reveal that deep learning (DL) models can detect and classify species using underwater fish images and obtain considerable results. “Fish-Dataset” is used for evaluations. This method corroborates significantly more discrimination accuracy ameliorations than the previously proposed techniques. The proposed model may be used for various underwater objects in light of the experimental findings.
Accurate Fish Detection under Marine Background Noise Based on the Retinex Enhancement Algorithm and CNN

Abstract:Underwater detection equipment with fish detection technology has broad application prospects in marine fishery resources exploration and conservation. In this paper, we establish a multi-scale retinex enhancement algorithm and a multi-scale feature-based fish detection model to improve underwater detection accuracy and ensure real-time performance. During image preprocessing, the enhancement algorithm combines the bionic structure of the fish retina and classical retinex theory to filter out underwater environmental noise. The detection model focuses on improving the detection performance on small-size targets using a deep learning method based on a convolutional neural network. We compare our method to current mainstream detection models (Faster R-CNN, RetinaNet, YOLO, SSDetc.), and the proposed model achieves better performance, with a mean Average Precision (mAP) of 78.31% and a mean Miss Rate (mMR) of 54.11% in the open fish image data set. The test results for the data from the field experiment prove the feasibility and stability of our model.
Computer vision in aquaculture: a case study of juvenile fish counting

Abstract:In aquaculture breeding or production programmes, counting juvenile fish represents a considerable cost in terms of the human hours needed. In this study, we explored the use of two state-of-the-art machine learning architectures (Single Shot Detection, hereafter SSD and Faster Regions with convolutional neural networks, hereafter Faster R-CNN) to augment a manual image-based juvenile fish counting method for the Australasian snapper (Chrysophrys auratus) bred at The New Zealand Institute for Plant and Food Research Limited. We tested model accuracy after tuning for confidence thresholds and non-maximal suppression overlap parameters, and implementing a bias correction using a Poisson regression model. Validation of image data showed that after tuning, bias-corrected SSD and Faster R-CNN models had mean absolute percent errors (MAPE) of less than 10%, with SSD having MAPE of less than 5%. Comparison of the results with those from manual counts showed that, while manual counts are slightly more accurate (MAPE = 1.56), the machine learning methods allow for more rapid assessment of counts and thus facilitating a higher throughput. This work represents a first step for deploying machine learning applications to an existing real-life aquaculture scenario and provides a useful starting point for further developments, such as real-time counting of fish or collecting additional phenotypic data from the source images.
Multi-class Fish Stock Statistics Technology Based on Object Classification and Tracking Algorithm

Abstract:The development of intensive aquaculture has increased the need for video-based underwater monitoring technology to generate statistics on multi-class fish. However, the complex marine environment, e.g., light fluctuations, shape deformations, similar appearance of fish, and occlusions, makes this a challenging task. Therefore, there are relatively few studies in this field. This paper proposes a real-time multi-class fish stock statistics method (RMCF). The accuracy of fish stock statistics has reached 95.6% over the previous best approach. The proposed method uses YOLOv4 as a backbone network and a parallel two-branch structure based on deep learning to perform real-time detection and tracking of fish in a real marine ranch environment. The two-branch structure contains detection and tracking branches, where the detection branch detects fish species and improves tracking accuracy and online tracking time. The tracking branch tracks the fish and making a number statistics. Finally, we combine the detection and tracking branches to generate multi-class fish stock statistics. Here, the detection branch helps the tracking branch realize multi-class tracking. With the tracking results, we further analyze the changing trends of different fish over time. Compared to state-of-the-art video tracking and detection methods, the experiment results demonstrate the proposed method provides better fish detection and tracking performance in a complex real-world marine environment.

Abstract:Intelligence technologies play an important role in increasing product quality and production efficiency in digital aquaculture. Automatic fish detection will contribute to achieving intelligent production and scientific management in precision farming. Due to the availability and ubiquity of modern information technology, such as the internet of things, big data, and camera devices, computer vision techniques, as an essential branch of artificial intelligence, have emerged as a powerful tool for achieving automatic fish detection. At present, it has been widely used in fish species identification, counting, and behavior analysis. Nevertheless, computer vision modeling used for fish detection is riddled with many challenges, such as varies in illumination, low contrast, high noise, fish deformation, frequent occlusion, and dynamic background. Hence, this paper provides a comprehensive review of the computer vision model for fish detection under unique application scenarios. Firstly, the image acquisition system based on 2D and 3D is discussed. Further, many fish detection techniques are categorized as appearance-based, motion-based, and deep learning. In addition, applications of fish detection and public open-source datasets are also presented in the literature. Finally, the prominent findings and the directions of future research are addressed toward the advancement in the aquaculture field throughout the discussion and conclusion section.

Abstract:<p>Fish behavior has attracted increasing attention in global aquaculture because it provides important information about productivity and fish quality. The use of images to detect fish behavior has shown potential in aquaculture behavioral studies by providing higher spatial resolution, efficiency, and accuracy than conventional approaches such as manual measurement. In addition, it allows for more quantitative data analysis than do other methods. To date, conventional image processing approaches to monitor fish behavior have been based primarily on appearance, morphology, and color information. This approach is complex and/or time-consuming and limits the practicality of such methods in aquaculture. To address these problems, we present herein a noninvasive, rapid, low-cost procedure based on an underwater imaging system and a deep learning framework to detect fish behavior with high accuracy in a mixed polyculture system. The specific objectives of this study are (1) to design a low-cost underwater imaging system that can describe and quantify fish behavior via visual images, and (2) to develop a lightweight deep learning structure to rapidly and accurately detect fish behavior under various conditions. Toward this end, images of fish are first captured via a low-cost imaging system, following which they are preprocessed to reduce noise and enhance data information. Finally, an improved You Only Look Once version 3 Lite (YOLOv3-Lite) network with a novel backbone structure is used to improve the pooling block and loss function and thereby better recognize fish behavior. The proposed method was tested on a real dataset and produced a Precision of 0.897, a Recall of 0.884, an intersection over union of 0.892, and 240 frames per second. Furthermore, when compared with faster region-convolutional neural network, YOLO, YOLOv2, YOLOv3, and single shot multi-Box detector, the performance of each evaluation metric of the proposed method was improved by 10%–20%. This comprehensive analysis indicates that the proposed method provides state-of-the-art performance and may be used in fish farms.</p>

Abstract:Machine-assisted object detection and classification of fish species from Baited Remote Underwater Video Station (BRUVS) surveys using deep learning algorithms presents an opportunity for optimising analysis time and rapid reporting of marine ecosystem statuses. Training object detection algorithms for BRUVS analysis presents significant challenges: the model requires training datasets with bounding boxes already applied identifying the location of all fish individuals in a scene, and it requires training datasets identifying species with labels. In both cases, substantial volumes of data are required and this is currently a manual, labour-intensive process, resulting in a paucity of the labelled data currently required for training object detection models for species detection. Here, we present a "machine-assisted" approach for i) a generalised model to automate the application of bounding boxes to any underwater environment containing fish and ii) fish detection and classification to species identification level, up to 12 target species. A catch-all " fish " classification is applied to fish individuals that remain unidentified due to a lack of available training and validation data. Machine-assisted bounding box annotation was shown to detect and label fish on out-of-sample datasets with a recall between 0.70 and 0.89 and automated labelling of 12 targeted species with an F 1 score of 0.79. On average, 12% of fish were given a bounding box with species labels and 88% of fish were located and given a fish label and identified for manual labelling. Taking a combined, machine-assisted approach presents a significant advancement towards the applied use of deep learning for fish species detection in fish analysis and workflows and has potential for future fish ecologist uptake if integrated into video analysis software. Manual labelling and classification effort is still required, and a community effort to address the limitation presented by a severe paucity of training data would improve automation accuracy and encourage increased uptake.

Abstract:Acoustic cameras, or imaging sonars, are high-potential devices for many applications in aquatic ecology, notably for fisheries management and population monitoring. However, how to extract such data into high-value information without a time-consuming entire data set reading by an operator is still a challenge. Moreover, the analysis of acoustic imaging, due to its low signal-to-noise ratio, is a perfect training ground for experimenting with new approaches, especially concerning deep learning techniques. We present hereby a novel approach that takes advantage of both convolutional neural network (CNN) and classical computer vision (CV) techniques, able to detect fish passages in acoustic video streams. The pipeline pre-treats the acoustic images to localise the signals of interest and to improve the detection performances. The YOLOv3-based model was trained with fish data from multiple species recorded by the two most frequently used models of acoustic cameras, the DIDSON and ARIS, including species of high ecological interest, as Atlantic salmon or European eels. The pre-treatment of images greatly improves the model performance, increasing its F1-score from 0.52 to 0.69. The model we developed provides satisfying results detecting almost 80% of fish passages and minimising the false-positive rate. On a validation data set, 40 h of videos and around 1 800 fish passages, the efficiency increases with the fish sizes, notably reaching a recall higher than 95% for Atlantic salmon. Conversely, the model appears much less efficient for eel detections on ARIS videos than on DIDSON data (31% recall vs 75%).

Abstract:Assessing the health of fish populations relies on determining the length of fish in sample species subsets, in conjunction with other key ecosystem markers; thereby, inferring overall health of communities. Despite attempts to use artificial intelligence (AI) to measure fish, most measurement remains a manual process, often necessitating fish being removed from the water. Overcoming this limitation and potentially harmful intervention by measuring fish without disturbance in their natural habitat would greatly enhance and expedite the process. Stereo baited remote underwater video systems (stereo-BRUVS) are widely used as a non-invasive, stressless method for manually counting and measuring fish in aquaculture, fisheries and conservation management. However, the application of deep learning (DL) to stereo-BRUVS image processing is showing encouraging progress towards replacing the manual and labour-intensive task of precisely locating the heads and tails of fish with computer-vision-based algorithms. Here, we present a generalised, semi-automated method for measuring the length of fish using DL with near-human accuracy for numerous species of fish. Additionally, we combine the DL method with a highly precise stereo-BRUVS calibration method, which uses calibration cubes to ensure precision within a few millimetres in calculated lengths. In a human versus DL comparison of accuracy, we show that, although DL commonly slightly over-estimates or under-estimates length, with enough repeated measurements, the two values average and converge to the same length, demonstrated by a Pearson correlation coefficient (r) of 0.99 for n=3954 measurement in 'out-of-sample' test data. We demonstrate, through the inclusion of visual examples of stereo-BRUVS scenes, the accuracy of this approach. The head-to-tail measurement method presented here builds on, and advances, previously published object detection for stereo-BRUVS. Furthermore, by replacing the manual process of four careful mouse clicks on the screen to precisely locate the head and tail of a fish in two images, with two fast clicks anywhere on that fish in those two images, a significant reduction in image processing and analysis time is expected. By reducing analysis times, more images can be processed; thereby, increasing the amount of data available for environmental reporting and decision making.

Abstract:Accurate fish species identification is essential for stock assessments, production management, document ecosystem changes, and protection of endangered species. Image processing and computer vision techniques have been widely employed for fish species detection, classification, and tracking, reducing human efforts in these tasks. However, these methods often rely on extensive training data with correct annotations. Annotating many images captured from marine environments poses a significant challenge. This work proposes a deep-learning model designed for fish detection and classification. The model incorporates an attention mechanism named Convolutional Block Attention Module (CBAM) to improve detection performance. A popular Deep Active Learning approach with cost-efficient annotation is employed, which selects the most informative samples from the unlabeled set. The proposed method utilizes probabilistic modeling based on mixture density networks to estimate probability distributions for localization and classification heads. This study uses the Southeast Area Monitoring and Assessment Program Dataset 2021 (SEAMAPD21). Our model is compared with the conventional supervised algorithm. Experimental results demonstrate superior detection accuracy, achieving a mean average precision (mAP) of 41.6% with minimal labeled data, compared to traditional supervised approaches (mAP-36.7%) that rely on larger labeled datasets. The active learning method with the attention module effectively reduces annotation costs while maintaining excellent detection accuracy. Overall, our proposed deep active learning model with an attention mechanism proves to be highly effective for fish species recognition, providing significant advancements in accuracy and cost efficiency for fish detection tasks.

Abstract:The United Nations' Sustainable Development Goals (SDGs) underscore aquaculture as a sustainable practice. However, many countries rely on ineffective conventional methods to monitor the aquaculture. Fish behaviour monitoring systems lack an integrated strategy, often focusing on underwater footage analysis or water quality data. Additionally, limited research exists on using learning algorithms to identify sensor data anomalies, limiting the effectiveness of such systems. This study proposes a comprehensive and effective aquaculture monitoring system to address these issues. The work introduces a novel method integrating fish motion analysis with water quality metrics. The study also presents a learning system that anticipates potential water quality parameters. The proposed model has the potential to significantly enhance aquaculture management procedures and contribute to the UN's SDGs through its ability to forecast water quality parameters and detect abnormal behaviour without requiring training detection and tracking algorithms. The study employs a large aquarium to capture water quality parameters and fish movement patterns. The study develops an FPGA-based water quality monitoring system and a prediction model to forecast potential water quality metrics. Among multiple LSTM models, the bi-directional LSTM performs well, achieving an RMSE score of 1.01 for water quality prediction. Subsequently, an outlier detection system is applied to identify unusual water quality parameters, triggering the behaviour analysis model. The behaviour analysis model uses an auto-encoder-based reconstruction approach to detect the frantic patterns in fish. The suggested behaviour analysis model has a f1-score of 0.68, demonstrating its reliability in contrast to conventional methods. The developed system is also tested on aquaculture site videos and includes a novel dataset of Sillago sihama with annotations for frantic behaviour patterns. The system works effectively as a decision support system for aquaculture.

Abstract:This study seeks to enhance aquaculture and fishery management using artificial intelligence, focusing on Nigerian catfish farming. The methodology encompasses a sequence of steps from data collection to validation. A dataset, primarily composed of aerial imagery from catfish ponds and supplemented with additional data from the internet, formed the foundation of this research. By leveraging computer vision and deep learning techniques, the data were processed to assess the potential of the three distinct cutting-edge object detection models. Based on various evaluation metrics to gauge their effectiveness in fish detection tasks, the Faster R-CNN emerged as the optimal model, boasting a superior balance of precision and recall. This model was subsequently integrated with an object-tracking model and deployed as an application, yielding promising results in terms of fish detection and tracking. The findings in this study suggest that AI-driven tools can automate monitoring processes, significantly increasing accuracy and efficiency in resource utilization.

Abstract:With the burgeoning global demand for seafood, potential solutions like aquaculture are increasingly significant, provided they address issues like pollution and food security challenges in a sustainable manner. However, significant obstacles such as disease outbreaks and inaccurate biomass estimation underscore the need for optimized solutions. This paper proposes "Fish-Sense", a deep learning-based pipeline inspired by the human visual system's ability to recognize and classify objects, developed in conjunction with fish farms, aiming to enhance disease detection and biomass estimation in the aquaculture industry. Our automated framework is two-pronged: one module for biomass estimation using deep learning algorithms to segment fish, classify species, and estimate biomass; and another for disease symptom detection symptoms, employing deep learning algorithms to classify fish into healthy and unhealthy categories, and subsequently identifying symptoms and locations of bacterial infections if a fish is classified as unhealthy. To overcome data scarcity in this field, we have created four novel real-world datasets for fish segmentation, health classification, species classification, and fish part segmentation. Our biomass estimation algorithms demonstrated substantial accuracy across five species, and the health classification. These algorithms provide a foundation for the development of industrial software solutions to improve fish health monitoring in aquaculture farms. Our integrated pipeline facilitates the transition from research to real-world applications, potentially encouraging responsible aquaculture practices. Nevertheless, these advancements must be seen as part of a comprehensive strategy aimed at improving the aquaculture industry's sustainability and efficiency, in line with the United Nations' Sustainable Development Goals' evolving interpretations. Abstract:Unlike land, the oceans, although covering more than 70% of the planet, are largely unexplored. Global fisheries resources are central to the sustainability and quality of life on earth but are under threat from climate change, ocean acidification and over consumption. One way to analyze these marine resource is through remote underwater surveying. However, the sheer volume of recorded data often make classification and analyses difficult, time consuming and resource intensive. Recent developments in machine learning (ML) have shown promising application in extracting high level context with near human performance on image classification tasks. The application of ML in remote underwater surveying can drastically reduce the processing time of these datasets. In order to train these deep neural networks used in ML, it is necessary to create a series of large-scale benchmark datasets to test any proposed algorithm for this kind of specific imaging classification. Currently, none of the publicly available datasets in the marine vision research domain have sufficiently large data volumes to reliably train a deep model. In this work, a publicly available large-scale benchmark underwater video dataset is created and used to retrain a state-of-the-art machine vision deep model (MaskRCNN). This model is in turn applied into detecting and classifying underwater marine lives through random under-sampling (RUS), and achieves a reasonably high average precision (0.628 mAP), indicating great applicability of this dataset in training instance segmentation deep neural network for detecting underwater marine species.

Abstract:Dithiocarbamates (DDTC) are chemicals widely used in the form of pesticides, therapeutic and chelating agents, and scavengers. Since DDTC interfere with SH, Cu, and Zn enzymes due to chelating properties, it was of interest to clarify, in primary culture of type II alveolar pneumocytes, the effect of this compound upon enzymes of glutathione cycle, Cu, Zn-superoxide dismutase, and the membrane structure of cells. DDTC significantly inhibited the activity of superoxide dismutase and the activity of gamma-glutamyl transpeptidase, glutathione reductase, and alkaline phosphatase, whereas an increase in the activity of glutathione peroxidase was found. The membranes of pneumocytes type II were injured. Data show that DDTC adversely affected type II pneumocyte function and structure.

Abstract:Monitoring an ornamental fish farm, like controlling the fish pond, is very a difficult task for farmers, as farmers need to be present in the farm and have to go with manual procedures with the cost of time, effort, and money. In this technology-advanced world, every work is done in a time limit and effortless manner. This paper suggests a system through which farmers can detect fish in underwater environment in any condition, like in turbid water or in dark environment. YOLOv5-CNN detection model is referred to as an advanced model for object detection and was used for this study, as it is better than the R-CNN model with respect to speed and accuracy. The images were trained using Labelimg, and the coding process was performed in Google Colab. The model was able to detect fish in real time with a probability score. The accuracy (mean average precision) of the model was 0.86. The model was tested with both images and videos; it was a promising result regarding the detection of fish in underwater environment.

Abstract:Inspired by the ambitions envisioned in the Fourth Industrial Revolution for aquaculture, also known as Aquaculture 4.0, the aquaculture (marine animal farming) industry is seeking to adopt data-driven Artificial Intelligence (AI) to help significantly improve business operations. One of the major barriers is the manual annotation of animal behaviour data, which is a time-consuming task that demands high levels of concentration from biologists. To address this challenge, this paper proposes novel automatic animal behaviour monitoring tailored for industrial scenarios. Our approach introduces a real-time machine-learning-based instance segmentation system that is specialised for underwater environments, where large groups of shrimp are farmed. The implemented system achieves an accuracy rate of 89% at 30 frames per second (fps) and can accurately detect shrimp in high-density areas under poor lighting conditions and high turbidity waters, despite the challenges of occlusion and overlapping. A key innovation of our method is the implementation of a new density cluster algorithm for time series and video analysis. This approach provides a more efficient and accurate way of monitoring animal behaviour, significantly saving time and effort for biologists and advancing the capabilities of automated aquaculture systems.

Abstract:Uses of underwater videos to assess diversity and abundance of fish are being rapidly adopted by marine biologists. Manual processing of videos for quantification by human analysts is time and labour intensive. Automatic processing of videos can be employed to achieve the objectives in a cost and time-efficient way. The aim is to build an accurate and reliable fish detection and recognition system, which is important for an autonomous robotic platform. However, there are many challenges involved in this task (e.g. complex background, deformation, low resolution and light propagation). Recent advancement in the deep neural network has led to the development of object detection and recognition in real time scenarios. An end-to-end deep learning-based architecture is introduced which outperformed the state of the art methods and first of its kind on fish assessment task. A Region Proposal Network (RPN) introduced by an object detector termed as Faster R-CNN was combined with three classification networks for detection and recognition of fish species obtained from Remote Underwater Video Stations (RUVS). An accuracy of 82.4% (mAP) obtained from the experiments are much higher than previously proposed methods.
A Deep Learning-Based Lightweight Model for the Detection of Marine Fishes

Abstract:The species and population size of marine fish are important for maintaining the ecological environment and reflecting climate change. Traditional fish detection methods mainly rely on manual or traditional computer vision, which has disadvantages such as complex design, low detection accuracy, and poor generalization. The widespread use of ocean observation systems has accumulated a large number of images and videos, which makes the application of deep learning on marine fish detection possible. In this paper, a real-time high-precision fish detection algorithm based on YOLOv5s is constructed. Considering the enhancement of the channel representation and spatial interaction ability of the model, the attention mechanism and gated convolution are introduced, respectively, and GhostNet is introduced to lighten the model. Through a series of model comparisons, two improved models, S-Head-Ghost-Fish9 and S-SE-HorBlock-Head-Ghost-Fish9, are finally obtained. Compared with the original model, in terms of model size, the former reduces by 19% and the latter increases by 9.5%; in terms of computation, the former reduces by 15.7% and the latter reduces by 3.1%; in terms of detection speed, both take about 17 ms to detect a single image, and both can meet the real-time detection requirements; in terms of detection accuracy, the former improves by 3% and the latter by 3.6%. Compared with the latest detection algorithms of YOLOv6 and YOLOv8, the detection accuracy is slightly lower than 1%, but the model size and computation amount are only 1/3 to 1/2 of them. The improved models can help assess the population size and growth of the fish, which is of great significance in maintaining the stability of the fish population.
Abnormal Behavior Monitoring Method of Larimichthys crocea in Recirculating Aquaculture System Based on Computer Vision

Abstract:It is crucial to monitor the status of aquaculture objects in recirculating aquaculture systems (RASs). Due to their high density and a high degree of intensification, aquaculture objects in such systems need to be monitored for a long time period to prevent losses caused by various factors. Object detection algorithms are gradually being used in the aquaculture industry, but it is difficult to achieve good results for scenes with high density and complex environments. This paper proposes a monitoring method for Larimichthys crocea in a RAS, which includes the detection and tracking of abnormal behavior. The improved YOLOX-S is used to detect Larimichthys crocea with abnormal behavior in real time. Aiming to solve the problems of stacking, deformation, occlusion, and too-small objects in a fishpond, the object detection algorithm used is improved by modifying the CSP module, adding coordinate attention, and modifying the part of the structure of the neck. After improvement, the AP50 reaches 98.4% and AP50:95 is also 16.2% higher than the original algorithm. In terms of tracking, due to the similarity in the fish's appearance, Bytetrack is used to track the detected objects, avoiding the ID switching caused by re-identification using appearance features. In the actual RAS environment, both MOTA and IDF1 can reach more than 95% under the premise of fully meeting real-time tracking, and the ID of the tracked Larimichthys crocea with abnormal behavior can be maintained stably. Our work can identify and track the abnormal behavior of fish efficiently, and this will provide data support for subsequent automatic treatment, thus avoiding loss expansion and improving the production efficiency of RASs.
