Abstract:Semantic segmentation suffers from the contradiction between inference speed and model accuracy. State-of-the-art real-time methods improve inference rapidity by sacrificing feature representation and model capacity. This paper proposes a novel Efficient Hybrid Attention Network (EHANet) to remedy this dilemma. The EHANet follows an encoder-decoder structure, where the encoder is composed of Reduced Basic-Block (RBB) with very few parameters. At decoding stages, a hybrid attention mechanism is designed to re-weight the feature map. The attention mechanism employs contextual attention for deep features and spatial attention for shallow features. The proposed architecture makes a trade off between inference speed and segmentation performance. As a result, the proposed model achieves 66.1% mIoU on the Cityscapes validation set. Meanwhile, it can operate at a speed of 113 FPS on one NVIDIA Titan XP GPU for an input image with size of 1024×512.

Abstract:The fusion of multi-scale features has been an effective method to get state-of-the-art performance in semantic segmentation. In this work, we concentrate on two tricky problems—the intra-class inconsistency and the blur on the localization of object boundaries and tackle them by combining two separate multi-scale context features respectively. Specifically, we propose a dual-stream structure with the scale context selection attention module to enhance the capabilities for multi-scale processing, where one stream collects global-scale context and the other captures local-scale information. Meanwhile, the embedded scale context selection attention module in each stream can adaptively focus on different scale context information to get optimal scale features. Based on our dual-stream structure with attention modules, our network can efficiently make use of multi-scale context to generate more comprehensive and powerful features. Our experiments show that our dual-stream network with scale context selection attention module achieves promising performance on the PASCAL VOC 2012 and PASCAL-Person-Part datasets.

Abstract:Abstract Currently, many real-time semantic segmentation networks aim for heightened accuracy, inevitably leading to increased computational complexity and reduced inference speed. Therefore, striking a balance between accuracy and speed has emerged as a crucial concern in this domain. To address these challenges, this study proposes a dual-branch fusion network with multiscale atrous pyramid pooling aggregate contextual features for real-time semantic segmentation (MAFNet). The first key component, the semantics guide spatial-details module (SGSDM) not only facilitates precise boundary extraction and fine-grained classification, but also provides semantic-based feature representation, thereby enhancing support for spatial analysis and decision boundaries. The second component, the multiscale atrous pyramid pooling module (MSAPPM), is designed by combining dilation convolution with feature pyramid pooling operations at various dilation rates. This design not only expands the receptive field, but also aggregates rich contextual information more effectively. To further improve the fusion of feature information generated by the dual-branch, a bilateral fusion module (BFM) is introduced. This module employs cross-fusion by calculating weights generated by the dual-branch to balance the weight relationship between the dual branches, thereby achieving effective feature information fusion. To validate the effectiveness of the proposed network, experiments are conducted on a single A100 GPU. MAFNet achieves a mean intersection over union (mIoU) of 77.4% at 70.9 FPS on the Cityscapes test dataset and 77.6% mIoU at 192.5 FPS on the CamVid test dataset. The experimental results conclusively demonstrated that MAFNet effectively strikes a balance between accuracy and speed.

Abstract:Semantic segmentation has made notable strides in analysing homogeneous large-scale 3D scenes, yet its application to varied scenes with diverse characteristics poses considerable challenges. Traditional methods have been hampered by the dependence on resource-intensive neighborhood search algorithms, leading to elevated computational demands. To overcome these limitations, we introduce the MFAF-SCNet, a novel and computationally streamlined approach for voxel-based sparse convolutional. Our key innovation is the multi-scale feature adaptive fusion (MFAF) module, which intelligently applies a spectrum of convolution kernel sizes at the network’s entry point, enabling the extraction of multi-scale features. It adaptively calibrates the feature weighting to achieve optimal scale representation for different objects. Further augmenting our methodology is the LKSNet, an original sparse convolutional backbone designed to tackle the inherent inconsistencies in point cloud distribution. This is achieved by integrating inverted bottleneck structures with large kernel convolutions, significantly bolstering the network’s feature extraction and spatial correlation proficiency. The efficacy of MFAF-SCNet was rigorously tested against three large-scale benchmark datasets—ScanNet and S3DIS for indoor scenes, and SemanticKITTI for outdoor scenes. The experimental results underscore our method’s competitive edge, achieving high-performance benchmarks while ensuring computational efficiency.

Abstract:Real-time semantic segmentation is a crucial technology in automatic driving scenarios, which needs to meet both high precision and real-time. The authors observe that learning complex correlations between object categories is vital in the real-time semantic segmentation task. Moreover, image spatial detail information plays an important role in small object segmentation and preserving edges and textures. A Semantics Recalibration and Detail Enhancement Network for real-time semantic segmentation based on BiSeNet V2 is proposed. On the one hand, a lightweight Semantics Recalibration module is designed to effectively extract global semantic contextual information, which combines pyramid segmentation and adaptive recalibration operations to learn the correlations between object categories. On the other hand, a Detail Enhancement module takes the feature maps of the shallow layers in the semantics branch as input and refines the feature maps to highlight the detail information. Finally, quantitative and qualitative analyses on Cityscapes and CamVid datasets demonstrate the effectiveness and generalisation of the proposed method.

Abstract:Semantic segmentation requires both rich spatial information and sizeable receptive field. However, modern approaches usually compromise spatial resolution to achieve real-time inference speed, which leads to poor performance. In this paper, we address this dilemma with a novel Bilateral Segmentation Network (BiSeNet). We first design a Spatial Path with a small stride to preserve the spatial information and generate high-resolution features. Meanwhile, a Context Path with a fast downsampling strategy is employed to obtain sufficient receptive field. On top of the two paths, we introduce a new Feature Fusion Module to combine features efficiently. The proposed architecture makes a right balance between the speed and segmentation performance on Cityscapes, CamVid, and COCO-Stuff datasets. Specifically, for a 2048x1024 input, we achieve 68.4% Mean IOU on the Cityscapes test dataset with speed of 105 FPS on one NVIDIA Titan XP card, which is significantly faster than the existing methods with comparable performance.

Abstract:Existing semantic segmentation networks perform well in accuracy by spending much computation. However, for practical applications, not only high segmentation accuracy but also high inference speed is required. To solve the problem of the difficult balance between accuracy and speed, we propose a new real-time semantic segmentation network (FBRNet). To extract multi-scale semantic information more quickly, we propose a lightly weighted reinforced atrous spatial pyramid pooling module (arASPP) based on the attention mechanism, which can extract richer and more advanced features with less computation than the original ASPP. To eliminate the semantic gap between high- and low-level features, we propose a new feature fusion module (CSFM), in which a shuffling mechanism is introduced to enhance robustness, and a parallel contextual information enhancement module and detail information enhancement module are built to facilitate the information exchange between high- and low-level features, achieving the effect of improving the model feature representation. Finally, we also introduce high-level features, fusing Laplace convolution and spatial attention mechanisms, and design the edge feature reinforcement module (LABRM) to eliminate the noise of low-level features and compensate for the model's segmentation effect target boundary. In the Cityscapes validation set and test set, FBRNet achieves 77.63% and 75.3% mIoU, and 101.9 FPS on a single tesla-T4 GPU, also achieved 72.4% mIoU and 89.8 FPS on the CamVid dataset and 55.2% mIoU and 100.8 FPS on the BDD100K dataset, which is a better balance of accuracy and speed compared with existing networks. IMM-Net: Integrated Multi-stream Memory Network for Real-Time Semantic Segmentation

Abstract:Real-time semantic segmentation is a challenging topic in computer vision. The popular BiSeNet utilizes twobranch approach for spatial information and context information independently. However, we find that its additional, coarser downsampling path to encode spatial information may cause structure redundancy. In this paper, an efficient and effective Integrated Multi-stream Memory module is designed and seamlessly integrated into the whole network architecture (termed IMM-Net) to obtain an extensive range of receptive fields and efficiently integrate multi-scale contextual information. Considering spatial location information is essential to preserving object boundaries, a specific Feature Aggregation Guidance Module is proposed to encode both interpixel semantic relationships and long-range location relationships. Comprehensive experiments on Cityscapes and CamVid datasets indicate our IMM-Net outperforms a few state-of-the-art real-time semantic segmentation methods, achieving a good speed-accuracy trade-off.

Abstract:In recent years, how to strike a good trade-off between accuracy, inference speed, and model size has become the core issue for real-time semantic segmentation applications, which plays a vital role in real-world scenarios such as autonomous driving systems and drones. In this study, we devise a novel lightweight network using a multi-scale context fusion (MSCFNet) scheme, which explores an asymmetric encoder-decoder architecture to alleviate these problems. More specifically, the encoder adopts some developed efficient asymmetric residual (EAR) modules, which are composed of factorization depth-wise convolution and dilation convolution. Meanwhile, instead of complicated computation, simple deconvolution is applied in the decoder to further reduce the amount of parameters while still maintaining the high segmentation accuracy. Also, MSCFNet has branches with efficient attention modules from different stages of the network to well capture multi-scale contextual information. Then we combine them before the final classification to enhance the expression of the features and improve the segmentation efficiency. Comprehensive experiments on challenging datasets have demonstrated that the proposed MSCFNet, which contains only 1.15M parameters, achieves 71.9% Mean IoU on the Cityscapes testing dataset and can run at over 50 FPS on a single Titan XP GPU configuration.

Abstract:Low-level details and high-level semantics are both essential to the semantic segmentation task. However, to speed up the model inference, current approaches almost always sacrifice the low-level details, leading to a considerable decrease in accuracy. We propose to treat these spatial details and categorical semantics separately to achieve high accuracy and high efficiency for real-time semantic segmentation. For this purpose, we propose an efficient and effective architecture with a good trade-off between speed and accuracy, termed Bilateral Segmentation Network (BiSeNet V2). This architecture involves the following: (i) A detail branch, with wide channels and shallow layers to capture low-level details and generate high-resolution feature representation; (ii) A semantics branch, with narrow channels and deep layers to obtain high-level semantic context. The detail branch has wide channel dimensions and shallow layers, while the semantics branch has narrow channel dimensions and deep layers. Due to the reduction in the channel capacity and the use of a fast-downsampling strategy, the semantics branch is lightweight and can be implemented by any efficient model. We design a guided aggregation layer to enhance mutual connections and fuse both types of feature representation. Moreover, a booster training strategy is designed to improve the segmentation performance without any extra inference cost. Extensive quantitative and qualitative evaluations demonstrate that the proposed architecture shows favorable performance compared to several state-of-the-art real-time semantic segmentation approaches. Specifically, for a input, we achieve 72.6% Mean IoU on the Cityscapes test set with a speed of 156 FPS on one NVIDIA GeForce GTX 1080 Ti card, which is significantly faster than existing methods, yet we achieve better segmentation accuracy. Abstract:Lightweight semantic segmentation plays an essential role in image signal processing that is beneficial to many multimedia applications, such as self-driving, robotic vision, and virtual reality. Due to the powerful capability to encode image details and semantics, many lightweight dual-resolution networks have been proposed in recent years for semantic segmentation. In spite of achieving remarkable progresses, they often ignore semantic context ranged from different scales. Furthermore, most of them always neglect the object boundaries, serving as a significant assistance for lightweight semantic segmentation. To alleviate these problems, this paper develops a Boundary-guide dual-resolution lightweight network with multi-scale Semantic Context, called BSCNet, for semantic segmentation. Specifically, to enhance the capability of feature representation, an Extremely Lightweight Pyramid Pooling Module (ELPPM) is designed to capture multi-scale semantic context at the top of low-resolution branch of BSCNet. In addition, to increase feature similarity of the same object while keeping feature discrimination of different objects, pixel information is propagated throughout the entire object area using a simple Boundary Auxiliary Fusion Module (BAFM), where the predicted object boundaries are served as high-level guidance to refine low-level convolutional features. The comprehensive experimental results have demonstrated that our BSCNet is simple and effective, achieving state-of-the-art trade-off in terms of segmentation accuracy and running efficiency on CityScapes, CamVid, and KITTI datasets.

Abstract:In semantic segmentation, an input image is partitioned into multiple meaningful segments each corresponding to a specific object or region. Multi-scale context plays a vital role in the accurate recognition of objects of different sizes and hence is key to overall accuracy enhancement. To achieve this goal, we introduce a novel strategy called Distributed Multi-scale Pyramid Pooling (DMPP) to extract multi-scale context at multiple levels of feature hierarchy. More specifically, we employ Pyramid Pooling Modules (PPM) in a distributed fashion after all three stages during the encoding phase. This enhances the feature representation capability of the network and leads to better performance. To extract context at a more granular level, we propose an Efficient Multi-scale Context Aggregation (EMCA) module which uses a combination of small and large kernels with large and small dilation rates, respectively. This alleviates the problem of sparse sampling and leads to consistent recognition of different regions. Apart from model accuracy, small model size and efficient execution are critically important for real-time mobile applications. To achieve it, we employ a resource-friendly combination of depthwise and factorized convolutions in the EMCA module to drastically reduce the number of parameters without significantly compromising the accuracy. Based on the EMCA module and DMPP, we propose a lightweight and real-time Distributed Multi-scale Pyramid Network (DMPNet) that achieves an excellent accuracy-efficiency trade-off. We also conducted extensive experiments on both driving datasets (i.e., Cityscapes and CamVid) and a general-purpose dataset (i.e., ADE20K) to show the effectiveness of the proposed method.

Abstract:The convolutional neural network achieves excellent semantic segmentation results in artificially annotated datasets with complex scenes. However, semantic segmentation methods still suffer from several problems such as low use rate of the features, high computational complexity, and being far from practical real-time application, which bring about challenges for the image semantic segmentation. Two factors are very critical to semantic segmentation task: global context and multilevel semantics. However, generating these two factors will always lead to high complexity. In order to solve this, we propose a novel structure, dual attention fusion module (DAFM), by eliminating structural redundancy. Unlike most of the existing algorithms, we combine the attention mechanism with the depth pyramid pool module (DPPM) to extract accurate dense features for pixel labeling rather than complex expansion convolution. Specifically, we introduce a DPPM to execute the spatial pyramid structure in output and combine the global pool method. The DAFM is introduced in each decoder layer. Finally, the low-level features and high-level features are fused to obtain semantic segmentation result. The experiments and visualization results on Cityscapes and CamVid datasets show that, in real-time semantic segmentation, we have achieved a satisfactory balance between accuracy and speed, which proves the effectiveness of the proposed algorithm. In particular, on a single 1080ti GPU computer, ResNet-18 produces 75.53% MIoU at 70 FPS on Cityscapes and 73.96% MIoU at 109 FPS on CamVid.

Abstract:In the realm of real-time semantic segmentation, deep neural networks have demonstrated promising potential. However, current methods face challenges when it comes to accurately segmenting object boundaries and small objects. This limitation is partly attributed to the prevalence of convolutional neural networks, which often involve multiple sequential down-sampling operations, resulting in the loss of fine-grained details. To overcome this drawback, we introduce BENet, a real-time semantic segmentation network with a focus on enhancing object boundaries. The proposed BENet integrates two key components: the boundary extraction module (BEM) and the boundary adaption layer (BAL). The proposed BEM efficiently extracts boundary information, while the BAL guides the network using this information to preserve intricate details during the feature extraction process. Furthermore, to address the challenges associated with poor segmentation of elongated objects, we introduce the strip mixed aggregation pyramid pooling module (SMAPPM). This module employs strip pooling kernels to effectively expand the contextual representation and receptive field of the network, thereby enhancing overall segmentation performance. Our experiments conducted on a single RTX 3090 GPU show that our method achieves an mIoU of 79.4% at a speed of 45.5 FPS on the Cityscapes test set without ImageNet pre-training.

MCFNet: Multi-scale Covariance Feature Fusion Network for Real-time Semantic Segmentation

Abstract:The low-level spatial detail information and high-level semantic abstract information are both essential to the semantic segmentation task. The features extracted by the deep network can obtain rich semantic information, while a lot of spatial information is lost. However, how to recover spatial detail information effectively and fuse it with high-level semantics has not been well addressed so far. In this paper, we propose a new architecture based on Bilateral Segmentation Network (BiseNet) called Multi-scale Covariance Feature Fusion Network (MCFNet). Specifically, this network introduces a new feature refinement module and a new feature fusion module. Furthermore, a gating unit named L-Gate is proposed to filter out invalid information and fuse multi-scale features. We evaluate our proposed model on Cityscapes, CamVid datasets and compare it with the state-of-the-art methods. Extensive experiments show that our method achieves competitive success. On Cityscapes, we achieve 75.5% mIOU with a speed of 151.3 FPS.

Abstract:With the swift progress of deep learning and its wide application in semantic segmentation, the effect of semantic segmentation has been significantly improved. However, how to achieve a reasonable compromise between accuracy, model size, and inference speed is crucial. In this paper, we propose a lightweight multi-scale asymmetric encoder–decoder network (LMANet) that is designed on the basis of an encoder–decoder structure. First, an optimized bottleneck module is used to extract features from different levels, and different receptive fields are applied to obtain effective information on different scales. Then, a channel-attention module and a feature-extraction module are introduced to constitute the residual structure, and different feature maps are connected by a feature-fusion module to effectively improve segmentation accuracy. Finally, a lightweight multi-scale decoder is designed to recover the image, and a spatial attention module is added to recover the spatial details effectively. This paper has verified the proposed method on the Cityscapes dataset and CamVid dataset and achieved mean intersection over union (mIoU) of 73.9% and 71.3% with the inference speeds of 111 FPS and 118 FPS, respectively, and the number of parameters is only 0.85 M.

A Deep Semantic Segmentation Network with Semantic and Contextual Refinements

Abstract:Semantic segmentation is a fundamental task in multimedia processing, which can be used for analyzing, understanding, editing contents of images and videos, among others. To accelerate the analysis of multimedia data, existing segmentation researches tend to extract semantic information by progressively reducing the spatial resolutions of feature maps. However, this approach introduces a misalignment problem when restoring the resolution of high-level feature maps. In this paper, we design a Semantic Refinement Module (SRM) to address this issue within the segmentation network. Specifically, SRM is designed to learn a transformation offset for each pixel in the upsampled feature maps, guided by high-resolution feature maps and neighboring offsets. By applying these offsets to the upsampled feature maps, SRM enhances the semantic representation of the segmentation network, particularly for pixels around object boundaries. Furthermore, a Contextual Refinement Module (CRM) is presented to capture global context information across both spatial and channel dimensions. To balance dimensions between channel and space, we aggregate the semantic maps from all four stages of the backbone to enrich channel context information. The efficacy of these proposed modules is validated on three widely used datasets-Cityscapes, Bdd100K, and ADE20K-demonstrating superior performance compared to state-of-the-art methods. Additionally, this paper extends these modules to a lightweight segmentation network, achieving an mIoU of 82.5% on the Cityscapes validation set with only 137.9 GFLOPs.

Abstract:Aiming to provide solutions for problems proposed by the inaccurate segmentation of long objects and information loss of small objects in real-time semantic segmentation algorithms, this paper proposes a lightweight multi-branch real-time semantic segmentation network based on BiseNetV2. The new auxiliary branch makes full use of spatial details and context information to cover the long object in the field of view. Meanwhile, in order to ensure the inference speed of the model, the asymmetric convolution is used in each stage of the auxiliary branch to design a structure with low computational complexity. In the multi-branch fusion stage, the alignment-and-fusion module is designed to provide guidance information for deep and shallow feature mapping, so as to make up for the problem of feature misalignment in the fusion of information at different scales, and thus reduce the loss of small target information. In order to further improve the model's awareness of key information, a global context module is designed to capture the most important features in the input data. The proposed network uses an NVIDIA GeForce RTX 3080 Laptop GPU experiment on the road street view Cityscapes and CamVid datasets, with the average simultaneously occurring ratios reaching 77.1% and 77.4%, respectively, and the running speeds reaching 127 frames/s and 112 frames/s, respectively. The experimental results show that the proposed algorithm can achieve a real-time segmentation and improve the accuracy significantly, showing good semantic segmentation performance.
