Abstract:Background: Routine clinical factors play an important role in the clinical diagnosis of focal liver lesions (FLLs); however, they are rarely used in computer-assisted diagnosis. Therefore, we developed a deep learning (DL) radiomics model, and investigated its effectiveness in diagnosing FLLs using long-range contrast-enhanced ultrasound (CEUS) cines and clinical factors. Methods: Herein, 303 patients with pathologically confirmed FLLs after surgery at three hospitals were retrospectively enrolled and divided into a training cohort (n=203), internal validation (IV) cohort (n=50) from one hospital with the ratio of 4:1, and external validation (EV) cohort (n=50) from the other two hospitals. Four DL radiomics models, namely Four Stream 3D convolutional neural network (FS3D(U)) (trained with CEUS cines only), FS3DU*A (trained with CEUS tines and alpha fetoprotein), FS3D(U+H) (trained with CEUS tines and hepatitis), and FS3D(U+A+H) (trained with CEUS tines, alpha fetoprotein, and hepatitis), were formed based on 31) convolutional neural networks (CNNs). They used approximately 20-s preoperative CEUS tines and/or clinical factors to extract spatiotemporal features for the classification of FLLs and the location of the region of interest. The area under curve of the receiver operating characteristic and diagnosis speed were calculated to evaluate the models in the IV and EV cohorts, and they were compared with those of two radiologists. Two-sided belong tests were used to calculate the statistical differences between the models and radiologists. Results: FS3D(U+A+H), which incorporated CEUS tines, hepatitis, and alpha fetoprotein, achieved the highest area under curve of 0.969 (95% CI: 0.901-1.000) and 0.957 (95% CI: 0.894-1.000) among radiologists and other models in IV and EV cohorts, respectively. A significant difference was observed when comparing FS3D(U) and radiologist 2 (all P<0.05). The diagnosis speed of all the models was the same (10.76 s per patient), and it was two times faster than those of the radiologists (radiologist 1: 23.74 and 27.75 s; radiologist 2: 25.95 and 29.50 s in IV and EV cohorts, respectively). Conclusions: The proposed DL radiomics demonstrated excellent performance on the benign and malignant diagnosis of FLLs by combining CEUS cines and clinical factors. It could help the individualized characterization of FLLs, and enhance the accuracy of diagnosis in the future.

Abstract:Liver cancer is one of the leading causes of death worldwide. Computer-aided diagnoses play an important role in liver lesion diagnoses (classification). Recently, several deep-learning-based computer-aided diagnosis systems have been proposed for the classification of liver lesions. The effectiveness of these systems has been demonstrated; however, the main challenge in deep-learning-based medical image classification is the lack of annotated training samples. In this paper, we demonstrate that transfer learning and fine-tuning can significantly improve the accuracy of liver lesion classification, especially for small training samples. We used the residual convolutional neural network (ResNet), which is a state-of-the-art network, as our baseline network for focal liver lesion classification using multi-phase CT images. Fine-tuning significantly improved the classification accuracy from 83.7% to 91.2%. This classification accuracy (91.2%) is higher than that of state-of-the-art methods.
Combining Convolutional and Recurrent Neural Networks for Classification of Focal Liver Lesions in Multi-phase CT Images.

Abstract:Computer-aided diagnosis (CAD) systems are useful for assisting radiologists with clinical diagnoses by classifying focal liver lesions (FLLs) based on multi-phase computed tomography (CT) images. Although many studies have conducted in the field, there still remain two challenges. First, the temporal enhancement pattern is hard to represent effectively. Second, the local and global information of lesions both are necessary for this task. In this paper, we proposed a framework based on deep learning, called ResGL-BDLSTM, which combines a residual deep neural network (ResNet) with global and local pathways (ResGL Net) with a bi-directional long short-term memory (BDLSTM) model for the task of focal liver lesions classification in multi-phase CT images. In addition, we proposed a novel loss function to train the proposed framework. The loss function is composed of an inter-loss and intra-loss, which can improve the robustness of the framework. The proposed framework outperforms state-of-the-art approaches by achieving a 90.93% mean accuracy.
Deep Learning Method for Content-Based Retrieval of Focal Liver Lesions Using Multiphase Contrast-Enhanced Computer Tomography Images

Abstract:A content-based image retrieval (CBIR) system can support radiologists in making clinical diagnosis through image analysis. Multiphase contrast-enhanced computer tomography (CT) images are more effective than single contrast-enhanced CT images in detecting and characterizing focal liver lesions (FLLs). This study proposes a deep learning method for the CBIR of FLLs using multiphase contrast-enhanced CT images. We use deep convolutional neural networks (DCNNs) to extract the temporal– spatial features from multiphase CT images. Compared with the conventional low- and mid-level features, the high-level features extracted by the DCNN can significantly improve the retrieval accuracy. The effectiveness of the proposed method was demonstrated through experiments with our multiphase FLL CT dataset, which is called as MPCT-FLL dataset. The mean average precision (mAP) was improved from 0.76 to 0.84.

Abstract:Computer-aided diagnosis ( CAD) systems are useful in assisting radiologists with clinical diagnoses by classifying focal liver lesions based on computed tomography ( CT) images. Extracting discriminative features from CT images is a crucial step in CAD systems. Although deep neural networks have demonstrated immense success in the computer vision community, there still remain two challenges in this field of medical image analysis. First, there are only limited dataset. Second, the local and global information of lesions both are necessary for this task. In this study, inspired by the importance of global and local information, we propose a novel model for distinguishing diverse types of focal liver lesions, called residual CNN with global and local pathways ( ResNet-GL) model. The model uses both patches of lesion region ( local information) and a whole-lesion region ( global information) as inputs. Since the proposed ResNet-GL is a pixel-wise classification method ( it assigns a label to each pixel of the lesion), we used the normalized label map produced by the ResNet-GL as an input of support vector machines ( SVM) for classification of lesions. The effectiveness of our model is confirmed by the accuracy of our testing dataset, which is over 87%. Our results show that the proposed ResNet-GL model can not only achieves superior performance than state-of-the-art approaches, which are based on mid-level learning-based features, but also can achieve results better than other CNN-based approaches.
Deep Learning for Accurate Diagnosis of Liver Tumor Based on Magnetic Resonance Imaging and Clinical Data

Abstract:Background:Early-stage diagnosis and treatment can improve survival rates of liver cancer patients. Dynamic contrast-enhanced MRI provides the most comprehensive information for differential diagnosis of liver tumors. However, MRI diagnosis is affected by subjective experience, so deep learning may supply a new diagnostic strategy. We used convolutional neural networks (CNNs) to develop a deep learning system (DLS) to classify liver tumors based on enhanced MR images, unenhanced MR images, and clinical data including text and laboratory test results. Methods:Using data from 1,210 patients with liver tumors (N= 31,608 images), we trained CNNs to get seven-way classifiers, binary classifiers, and three-way malignancy-classifiers (Model A-Model G). Models were validated in an external independent extended cohort of 201 patients (N= 6,816 images). The area under receiver operating characteristic (ROC) curve (AUC) were compared across different models. We also compared the sensitivity and specificity of models with the performance of three experienced radiologists. Results:Deep learning achieves a performance on par with three experienced radiologists on classifying liver tumors in seven categories. Using only unenhanced images, CNN performs well in distinguishing malignant from benign liver tumors (AUC, 0.946; 95% CI 0.914-0.979 vs. 0.951; 0.919-0.982,P= 0.664). New CNN combining unenhanced images with clinical data greatly improved the performance of classifying malignancies as hepatocellular carcinoma (AUC, 0.985; 95% CI 0.960-1.000), metastatic tumors (0.998; 0.989-1.000), and other primary malignancies (0.963; 0.896-1.000), and the agreement with pathology was 91.9%.These models mined diagnostic information in unenhanced images and clinical data by deep-neural-network, which were different to previous methods that utilized enhanced images. The sensitivity and specificity of almost every category in these models reached the same high level compared to three experienced radiologists. Conclusion:Trained with data in various acquisition conditions, DLS that integrated these models could be used as an accurate and time-saving assisted-diagnostic strategy for liver tumors in clinical settings, even in the absence of contrast agents. DLS therefore has the potential to avoid contrast-related side effects and reduce economic costs associated with current standard MRI inspection practices for liver tumor patients.

Abstract:ObjectivesTo verify the value of deep learning in diagnosing nonalcoholic fatty liver disease (NAFLD) by comparing 3 image‐processing techniques. MethodsA total of 240 participants were recruited and divided into 4 groups (normal, mild, moderate, and severe NAFLD groups), according to the definition and the ultrasound scoring system for NAFLD. Two‐dimensional hepatic imaging was analyzed by the envelope signal, grayscale signal, and deep‐learning index obtained by 3 image‐processing techniques. The values of the 3 methods ranged from 0 to 65,535, 0 to 255, and 0 to 4, respectively. We compared the values among the 4 groups, draw receiver operating characteristic curves, and compared the area under the curve (AUC) values to identify the best image‐processing technique. ResultsThe envelope signal value, grayscale value, and deep‐learning index had a significant difference between groups and increased with the severity of NAFLD (P 0.7) to identify NAFLD. Meanwhile, the deep‐learning index showed the superior diagnostic ability in distinguishing moderate and severe NAFLD (AUC = 0.958). ConclusionsThe envelope signal and grayscale values were vital parameters in the diagnosis of NAFLD. Furthermore, deep learning had the best sensitivity and specificity in assessing the severity of NAFLD.

Abstract:Accurate analysis of the fibrosis stage plays very important roles in follow-up of patients with chronic hepatitis B infection. In this paper, a deep learning framework is presented for automatically liver fibrosis prediction. On contrary of previous works, our approach can take use of the information provided by multiple ultrasound images. An indicator-guided learning mechanism is further proposed to ease the training of the proposed model. This follows the workflow of clinical diagnosis and make the prediction procedure interpretable. To support the training, a dataset is well-collected which contains the ultrasound videos/images, indicators and labels of 229 patients. As demonstrated in the experimental results, our proposed model shows its effectiveness by achieving the state-of-the-art performance, specifically, the accuracy is 65.6%(20% higher than previous best).
Deep Learning-Assisted Diagnosis of Liver Tumors Using Non-Contrast Magnetic Resonance Imaging: A Multi-Center Study

Abstract:Background: Contrast-enhanced MRI is the best imaging modality for liver tumor detection and differential diagnosis. However, it is long scan times required and has the contrast agent-associated risks. This study aims to develop and validate a deep convolutional neural network for initial diagnosis of liver tumors based on non-contrast MRI. Methods: In total, 50418 images in enhanced MRI from 1959 patients with liver tumor in three center were enrolled. T2-weighted imaging, diffusion-weighted imaging (DWI), and multiphasic T1-weighted imaging provided input for Inception-ResNet V2 through transfer learning to generate four models for three-way classification. The models was then validated on the independent internal and two external datasets consisting of 5172 and 2916,1338 images, respectively. The diagnostic performance of non-contrast models(T2, T2+DWI) for distinguishing malignancy from benign tumors at-patient level were further evaluated in three validation sets. Findings: Non-contrast models demonstrated similar performance for classifying liver tumors to benign, primary malignant and metastatic tumors, compared with two models based on multi-sequence or enhanced images. In the independent internal cohort, the areas under the receiver operating characteristic curves of T2+DWI model reached 0.91(95% CI,0.888–0.932), 0.873(95% CI,0.848-0.899), and 0.876 (95% CI, 0.840-0.911) for three categories, respectively. At patient-level, the sensitivities of malignant tumors gained from non-contrast models reached 98.1%, 85.7%, 87.5% respectively in three validation sets, while all specificities were almost greater than 70%. Interpretation: This study demonstrates that based on non-contrast MRI, deep learning algorithm can correctly classify liver tumors into benign, primary malignant and metastatic tumors at image-level, and distinguish malignancy from benign with high sensitivity at patient-level, potentially reducing the number of enhanced testing to avoid side effects and financial costs. Abstract:Using ultrasound imaging to diagnose liver steatosis is of great significance for preventing diseases such as cirrhosis and liver cancer. Accurate diagnosis under conditions of low quality, noise and poor resolutions is still a challenging task. Physiological studies have shown that the visual cortex of the biological visual system has selective attention neural mechanisms and feedback regulation of high features to low features. When processing visual information, these cortical regions selectively focus on more sensitive information and ignore unimportant details, which can effectively extract important features from visual information. Inspired by this, we propose a new diagnostic network for hepatic steatosis. In order to simulate the selection mechanism and feedback regulation of the visual cortex in the ventral pathway, it consists of a receptive field feature extraction module, parallel attention module and feedback connection. The receptive field feature extraction module corresponds to the inhibition of the non-classical receptive field of V1 neurons on the classical receptive field. It processes the input image to suppress the unimportant background texture. Two types of attention are adopted in the parallel attention module to process the same visual information and extract different important features for fusion, which improves the overall performance of the model. In addition, we construct a new dataset of fatty liver ultrasound images and validate the proposed model on this dataset. The experimental results show that the network has good performance in terms of sensitivity, specificity and accuracy for the diagnosis of fatty liver disease.
Ultrasound‐Based Machine Learning Approach for Detection of Nonalcoholic Fatty Liver Disease

Abstract:Objectives Current diagnosis of nonalcoholic fatty liver disease (NAFLD) relies on biopsy or MR‐based fat quantification. This prospective study explored the use of ultrasound with artificial intelligence for the detection of NAFLD. Methods One hundred and twenty subjects with clinical suspicion of NAFLD and 10 healthy volunteers consented to participate in this institutional review board‐approved study. Subjects were categorized as NAFLD and non‐NAFLD according to MR proton density fat fraction (PDFF) findings. Ultrasound images from 10 different locations in the right and left hepatic lobes were collected following a standard protocol. MRI‐based liver fat quantification was used as the reference standard with >6.4% indicative of NAFLD. A supervised machine learning model was developed for assessment of NAFLD. To validate model performance, a balanced testing dataset of 24 subjects was used. Sensitivity, specificity, positive predictive value, negative predictive value, and overall accuracy with 95% confidence interval were calculated. Results A total of 1119 images from 106 participants was used for model development. The internal evaluation achieved an average precision of 0.941, recall of 88.2%, and precision of 89.0%. In the testing set AutoML achieved a sensitivity of 72.2% (63.1%–80.1%), specificity of 94.6% (88.7%–98.0%), positive predictive value (PPV) of 93.1% (86.0%–96.7%), negative predictive value of 77.3% (71.6%–82.1%), and accuracy of 83.4% (77.9%–88.0%). The average agreement for an individual subject was 92%. Conclusions An ultrasound‐based machine learning model for identification of NAFLD showed high specificity and PPV in this prospective trial. This approach may in the future be used as an inexpensive and noninvasive screening tool for identifying NAFLD in high‐risk patients.

Abstract:Background: The diagnosis performance of B-mode ultrasound (US) for focal liver lesions (FLLs) is relatively limited. We aimed to develop a deep convolutional neural network of US (DCNN-US) for aiding radiologists in classification of malignant from benign FLLs. Materials and methods: This study was conducted in 13 hospitals and finally 2143 patients with 24,343 US images were enrolled. Patients who had non-cystic FLLs with pathological results were enrolled. The FLLs from 11 hospitals were randomly divided into training and internal validations (IV) cohorts with a 4:1 ratio for developing and evaluating DCNN-US. Diagnostic performance of the model was verified using external validation (EV) cohort from another two hospitals. The diagnosis value of DCNN-US was compared with that of contrast enhanced computed tomography (CT)/magnetic resonance image (MRI) and 236 radiologists, respectively. Findings: The AUC of ModelLBC for FLLs was 0.924 (95% CI: 0.889–0.959) in the EV cohort. The diagnostic sensitivity and specificity of ModelLBC were superior to 15-year skilled radiologists (86.5% vs 76.1%, p = 0.0084 and 85.5% vs 76.9%, p = 0.0051, respectively). Accuracy of ModelLBC was comparable to that of contrast enhanced CT (both 84.7%) but inferior to contrast enhanced MRI (87.9%) for lesions detected by US. Interpretation: DCNN-US with high sensitivity and specificity in diagnosing FLLs shows its potential to assist less-experienced radiologists in improving their performance and lowering their dependence on sectional imaging in liver cancer diagnosis.

Abstract:Abstract Objective This study aims to develop a ResNet50‐based deep learning model for focal liver lesion (FLL) classification in ultrasound images, comparing its performance with other models and prior research. Methodology We retrospectively collected 581 ultrasound images from the Chulabhorn Hospital's HCC surveillance and screening project (2010–2018). The dataset comprised five classes: non‐FLL, hepatic cyst (Cyst), hemangioma (HMG), focal fatty sparing (FFS), and hepatocellular carcinoma (HCC). We conducted 5‐fold cross‐validation after random dataset partitioning, enhancing training data with data augmentation. Our models used modified pre‐trained ResNet50, GGN, ResNet18, and VGG16 architectures. Model performance, assessed via confusion matrices for sensitivity, specificity, and accuracy, was compared across models and with prior studies. Results ResNet50 outperformed other models, achieving a 5‐fold cross‐validation accuracy of 87 ± 2.2%. While VGG16 showed similar performance, it exhibited higher uncertainty. In the testing phase, the pretrained ResNet50 excelled in classifying non‐FLL, cysts, and FFS. To compare with other research, ResNet50 surpassed the prior methods like two‐layered feed‐forward neural networks (FFNN) and CNN+ReLU in FLL diagnosis. Conclusion ResNet50 exhibited good performance in FLL diagnosis, especially for HCC classification, suggesting its potential for developing computer‐aided FLL diagnosis. However, further refinement is required for HCC and HMG classification in future studies.

Abstract:The early detection of liver fibrosis is of significant importance. Deep learning analysis of ultrasound backscattered radiofrequency (RF) signals is emerging for tissue characterization as the RF signals carry abundant information related to tissue microstructures. However, the existing methods only used the time-domain information of the RF signals for liver fibrosis assessment, and the liver region of interest (ROI) is outlined manually. In this study, we proposed an approach for liver fibrosis assessment using deep learning models on ultrasound RF signals. The proposed method consisted of two-dimensional (2D) convolutional neural networks (CNNs) for automatic liver ROI segmentation from reconstructed B-mode ultrasound images and one-dimensional (1D) CNNs for liver fibrosis stage classification based on the frequency spectra (amplitude, phase, and power) of the segmented ROI signals. The Fourier transform was used to obtain the three kinds of frequency spectra. Two classical 2D CNNs were employed for liver ROI segmentation: U-Net and Attention U-Net. ROI spectrum signals were normalized and augmented using a sliding window technique. Ultrasound RF signals collected (with a 3-MHz transducer) from 613 participants (Group A) were included for liver ROI segmentation and those from 237 participants (Group B) for liver fibrosis stage classification, with a liver biopsy as the reference standard (Fibrosis stage: F0 = 27, F1 = 49, F2 = 51, F3 = 49, F4 = 61). In the test set of Group A, U-Net and Attention U-Net yielded Dice similarity coefficients of 95.05% and 94.68%, respectively. In the test set of Group B, the 1D CNN performed the best when using ROI phase spectrum signals to evaluate liver fibrosis stages ≥F1 (area under the receive operating characteristic curve, AUC: 0.957; accuracy: 89.19%; sensitivity: 85.17%; specificity: 93.75%), ≥F2 (AUC: 0.808; accuracy: 83.34%; sensitivity: 87.50%; specificity: 78.57%), and ≥F4 (AUC: 0.876; accuracy: 85.71%; sensitivity: 77.78%; specificity: 94.12%), and when using the power spectrum signals to evaluate ≥F3 (AUC: 0.729; accuracy: 77.14%; sensitivity: 77.27%; specificity: 76.92%). The experimental results demonstrated the feasibility of both the 2D and 1D CNNs in liver parenchyma detection and liver fibrosis characterization. The proposed methods have provided a new strategy for liver fibrosis assessment based on ultrasound RF signals, especially for early fibrosis detection. The findings of this study shed light on deep learning analysis of ultrasound RF signals in the frequency domain with automatic ROI segmentation.

Diagnosis of Cirrhosis Stage Via Deep Neural Network.

Abstract:This paper proposes a novel fully automatic diagnosis method for liver cirrhosis based on the reading of high-frequency ultrasound images. The proposed method determines the cirrhosis stage via a deep-learning neural network. First, we feed an ultrasound image into an autoencoder to generate the capsule-enhanced version of the image and binarize the enhanced image. Then, we employ a partition-clustering algorithm to obtain the top-end largest-area partition cluster, which represents the upper layer of the liver, and thereby locate the final liver capsule based on least-squares polynomial fitting. After separating the parenchymal region from the image, we use the proposed residual neural network to determine the cirrhosis stage. Experimental results demonstrate the high accuracy and effectiveness of the proposed method, which outperforms five other state-of-the-art methods. The proposed method is expected to improve the efficiency and accuracy of the clinical diagnosis of liver cirrhosis.

Abstract:Ultrasound imaging is a widely used technique for fatty liver diagnosis as it is practically affordable and can be quickly deployed by using suitable devices. When it is applied to a patient, multiple images of the targeted tissues are produced. We propose a machine learning model for fatty liver diagnosis from multiple ultrasound images. The machine learning model extracts features of the ultrasound images by using a pre-trained image encoder. It further produces a summary embedding on these features by using a graph neural network. The summary embedding is used as input for a classifier on fatty liver diagnosis. We train the machine learning model on a ultrasound image dataset collected by Taiwan Biobank. We also carry out risk control on the machine learning model using conformal prediction. Under the risk control procedure, the classifier can improve the results with high probabilistic guarantees.

Abstract:Non-alcoholic fatty liver disease (NAFLD) is a popular chronic disease worldwide, with a wide spectrum of conditions, ranging from fatty liver (NAFL) to non-alcoholic steatohepatitis (NASH). Liver biopsy is the gold standard to diagnose NAFLD. However, it is an invasive procedure that is prone to sampling error and can lead to complications, which makes it an urgent need to develop non-invasive tests. Ultrasound (US) is an inexpensive, nonionizing-radiative, and real-time imaging modality that is used widely in practice. Ballooning and inflammation are very important for evaluating NASH resolution. In this study, we stage ballooning and inflammation based on multi-modal US features extracted from radiofrequency (RF) data, B-mode images, shear wave elastography (SWE) images, and baseline data. The results demonstrated that the multi-modal quantitative US features can stage ballooning and inflammation with moderate or good performance, indicating that the multi-modal US features may be a promising way to guide liver biopsy and NASH resolution.

Abstract:Cirrhosis is a chronic liver disease that seriously jeopardizes the life and health of patients. Currently, ultrasound (US) imaging is commonly used by the computer-aided diagnosis (CAD) system to diagnose cirrhosis. With the rapid development of artificial intelligence, deep learning methods for cirrhosis diagnosis using ultrasound image data have emerged. However, due to US images’ complexity and variability, this input usually requires manual annotation. This study proposes LiverTL, an end-to-end deep learning approach for the automatic cirrhosis ultrasound image classification to overcome these limitations. LiverTL includes an automatic region of interest (ROI) detection module to support various ultrasound images’ ROI extraction. Simultaneously, the classification module utilizes ROI areas and obtain the cirrhosis diagnosis results through the transfer learning network. We find that LiverTL achieves high classification accuracy on our evaluation data set. The cirrhosis data experiments suggest that a proper pre-training model for transfer learning is crucial for the classification results. These findings potentially pave the way to advance the diagnosis and therapy of cirrhosis.
Automatic Detection and Classification of Focal Liver Lesions Based on Deep Convolutional Neural Networks: A Preliminary Study

Abstract:With the increasing daily workload of physicians, computer-aided diagnosis (CAD) systems based on deep learning play an increasingly important role in pattern recognition of diagnostic medical images. In this paper, we propose a framework based on hierarchical convolutional neural networks (CNNs) for automatic detection and classification of focal liver lesions (FLLs) in multi-phasic computed tomography (CT). A total of 616 nodules, composed of three types of malignant lesions (hepatocellular carcinoma, intrahepatic cholangiocarcinoma, and metastasis) and benign lesions (hemangioma, focal nodular hyperplasia, and cyst), were randomly divided into training and test sets at an approximate ratio of 3:1. To evaluate the performance of our model, other commonly adopted CNN models and two physicians were included for comparison. Our model achieved the best results to detect FLLs, with an average test precision of 82.8%, recall of 93.4%, and F1-score of 87.8%. Our model initially classified FLLs into malignant and benign and then classified them into more detailed classes. For the binary and six-class classification, our model achieved average accuracy results of 82.5 and73.4%, respectively, which were better than the other three classification neural networks. Interestingly, the classification performance of the model was placed between a junior physician and a senior physician. Overall, this preliminary study demonstrates that our proposed multi-modality and multi-scale CNN structure can locate and classify FLLs accurately in a limited dataset, and would help inexperienced physicians to reach a diagnosis in clinical practice.

Abstract:Liver fibrosis, inflammation and steatosis are three typical pathological forms of chronic liver diseases (CLDs) and affect lots of people worldwide. The early diagnosis and accurate grading of these three diseases are decisive for controlling the development of the diseases, promoting the reversal of the disease course and improving the prognosis of patients with CLDs. This study proposes an intelligent grading framework for these three diseases based on a multi-parametric quantitative ultrasound (QUS) method to extract both explicable handcrafted and high-dimensional deep features from multimodal ultrasound data, including B-mode images, shear wave elasticity (SWE) images and radio-frequency and envelope signals of transient elastography (TE). The handcrafted and deep features are fused and used as inputs of an artificial neural network (ANN) to grade liver fibrosis, inflammation and steatosis simultaneously. With accuracy (ACC), sensitivity (SEN), specificity (SPE) and area under the receiver operating characteristic curve (AUC) as the evaluation indexes, the proposed method performs well with all the evaluation indexes for all the three diseases higher than 0.82 and those for liver fibrosis higher than 0.84. The results show that the proposed method may be a promising and competitive tool for the intelligent diagnosis of the three typical pathological forms of CLDs.
