Abstract:Non-intrusive load monitoring (NILM) is a promising technique for energy consumption monitoring that can recognize load states and appliance types without relying on excessive sensing meters. With the development of the Internet of Things in intelligent buildings, the NILM technique will have broad application prospects. According to the different characteristics of load electrical signals, this work constructs 2D load signatures, including building the weighted voltage-current (WVI ) trajectory image, Markov Transition Field (MTF) image, and current spectral sequence-based GAF (I-GAF) image. Furthermore, a deep learning model named Residual Convolutional Neural Network with Energy-normalization and Squeeze-and-excitation blocks (EN-SE-RECNN) is proposed to mine information on the constructed load signatures and realize the appliance identification task. The accuracy of the proposed method on PLAID, WHITED, and HRAD datasets reached 97.43%, 95.99%, and 98.14%, respectively. And it shows that the proposed method significantly improves the recognition performance compared to existing methods. (c) 2022 Elsevier B.V. All rights reserved.

Abstract:Nonintrusive load monitoring (NILM) is a cost-effective technology for monitoring detailed electricity energy consumption. In recent years, machine learning has emerged as the predominant approach for achieving NILM tasks. However, machine learning models require an extensive volume of labeled data which is unachievable in the real world. Additionally, the collected power data is susceptible to noise interference arising from grid or measurement error. To this end, this article presents a new NILM method, adaptive variational mode extraction-Hilbert transform-excitation attention-semisupervised curriculum label learning (AVME-HT-EA-SCLL), which offers robust antinoise performance, comprehensive feature extraction, efficient utilization of unlabeled data, and exceptional classification accuracy. The main contributions of this work include the proposed adaptive variational mode extraction (AVME) method for efficient signal decomposition, a new feature extraction method, which combines AVME and Hilbert transform to extract unique features and filter out noise interference, a semisupervised learning (SSL) model based on curriculum learning strategy to identify appliances with limited labeled data, and an excitation attention (EA) network to amplify attention toward crucial information. Experimental evaluations conducted on public datasets such as the plug-load appliance identification dataset (PLAID) and the worldwide household and industry transient energy dataset (WHITED), as well as a private dataset collected in the laboratory, demonstrate that the proposed method surpasses state-of-the-art approaches.

Abstract:Deep learning models for non-intrusive load monitoring (NILM) tend to require a large amount of labeled data for training. However, it is difficult to generalize the trained models to unseen sites due to different load characteristics and operating patterns of appliances between data sets. For addressing such problems, self-supervised learning (SSL) is proposed in this paper, where labeled appliance-level data from the target data set or house is not required. Initially, only the aggregate power readings from target data set are required to pre-train a general network via a self-supervised pretext task to map aggregate power sequences to derived representatives. Then, supervised downstream tasks are carried out for each appliance category to fine-tune the pre-trained network, where the features learned in the pretext task are transferred. Utilizing labeled source data sets enables the downstream tasks to learn how each load is disaggregated, by mapping the aggregate to labels. Finally, the fine-tuned network is applied to load disaggregation for the target sites. For validation, multiple experimental cases are designed based on three publicly accessible REDD, UK-DALE, and REFIT data sets. Besides, state-of-the-art neural networks are employed to perform NILM task in the experiments. Based on the NILM results in various cases, SSL generally outperforms zero-shot learning in improving load disaggregation performance without any sub-metering data from the target data sets.

Abstract:Nonintrusive load monitoring (NILM) identifies the status and power consumption of various household appliances by disaggregating the total power usage signal of an entire house. Efficient and accurate load monitoring facilitates user profile establishment, intelligent household energy management, and peak load shifting. This is beneficial for both the end users and utilities by improving the overall efficiency of a power distribution network. Existing approaches mainly focus on developing an individual model for each appliance. Those approaches typically rely on a large amount of household-labeled data that are hard to collect. In this article, we propose a multi-appliance-task framework with a training-efficient sample augmentation (SA) scheme that boosts the disaggregation performance with limited labeled data. For each appliance, we develop a shared-hierarchical split structure for its regression and classification tasks. In addition, we also propose a 2-D attention mechanism in order to capture spatio-temporal correlations among all appliances. With only one-day training data and limited appliance operation profiles, the proposed SA algorithm can achieve comparable test performance to the case of training with the full dataset. Finally, simulation results show that our proposed approach features a significantly improved performance over many baseline models. The relative errors can be reduced by more than 50% on average.

Abstract:Awareness of electric energy usage has both societal and economic benefits, which include reduced energy bills and stress on non-renewable energy sources. In recent years, there has been a surge in interest in the field of load monitoring, also referred to as energy disaggregation, which involves methods and techniques for monitoring electric energy usage and providing appropriate feedback on usage patterns to homeowners. The use of unsupervised learning in non-intrusive load monitoring (NILM) is a key area of study, with practical solutions having wide implications for energy monitoring. In this paper, a low-complexity unsupervised NILM algorithm is presented, which is designed toward practical implementation. The algorithm is inspired by a fuzzy clustering algorithm called entropy index constraints competitive agglomeration, but facilitated and improved in a practical load monitoring environment to produce a set of generalized appliance models for the detection of appliance usage within a household. Experimental evaluation conducted using energy data from the reference energy data disaggregation dataset indicates that the algorithm has out-performance for event detection compared with recent state-of-the-art work for unsupervised NILM when considering common NILM metrics, such as accuracy, precision, recall, ${F}$ -measure, and total energy correctly assigned.

Abstract:Non-Intrusive Load Monitoring (NILM) increases awareness on user energy usage patterns. In this paper, an efficient and highly accurate NILM method is proposed featuring condensed representation, super-state and fusion of two deep learning based models. Condensed representation helps the two models perform more efficiently and preserve longer-term information, while super-state helps the model to learn correlations between appliances. The first model is a deep user model that learns user appliances usage patterns to predict the next appliance usage behavior based on past behaviors by capturing the dynamics of user behaviors history and appliances usage habits. The second model is a deep appliance group model that learns the characteristics of appliances with temporal and electrical information. These two models are then fused to perform NILM. The case study based on REFIT datasets demonstrates that the proposed NILM method outperforms two state-of-the-art benchmark methods.

Abstract:Non-Intrusive Load Monitoring (NILM) has become a research boom due to its energy-saving benefits as the smart grid develops and the greenhouse effect intensifies. However, existing NILM models may perform poorly in the target domains collected from different sources, or those containing unseen appliance types, blocking the rollout of NILM. In contrast to the methods that up-date the trained model on the unseen data to handle domain shift or heterogeneous label space, this paper proposes a novel general-izable NILM method based on metric-based meta-learning and su-pervised pre-training. It beforehand learns the cross-domain meta-knowledge through meta-training to eliminate the need for parameter updates in the target domain. Moreover, this method is specifically designed for practical deployments at the edge where both labeled instances and computation resources are limited. The proposed method transforms the appliance current into a metric vector via lightweight 1D convolution and then uses the relation module to propagate the labels via similarity. The experimental results on three public datasets and the proposed dataset demon-strate that the proposed method can achieve high generalization performance in different datasets, users houses, appliance brands, and appliance types.

Abstract:Non-Intrusive Load Monitoring (NILM) is particularly important for demand response. This paper proposes an innovative method based on a deep learning model to recognize the working state of electrical appliances using low frequency load data. The approach includes a data processing step, a deep learning model and a new accuracy calculation method. The data processing step consists of a multi-feature and high-dimensional method (MFHDM) and a pre-training process. The deep learning model consists of a convolutional neural network (CNN), a long-term short-term memory network (LSTM) and a random-forest (RF) algorithm. The proposed method addresses the label correlation problem and the class-imbalance problem. To test the proposed method, the Reference Energy Disaggregation Dataset (REDD) and the Pecan Street dataset (PSD) are used. A comparative analysis with several models shows that the proposed method can effectively improve electrical appliance recognition accuracy and realize NILM.

Abstract:The essence of Non-Intrusive Load Monitoring (NILM) is to extract electricity consumption details of individual appliance from an aggregated house-level electrical measurement at the main panel without sub-metering each appliance. In this paper, an Expectation Maximization (EM) based semi-supervised multi-label classification technique is applied in NILM. It requires a one-time registration of individual appliance to obtain few samples during the training stage. After that, the total electricity is utilized to detect the states of each appliance and analyze electricity consumption information of individual appliance for each instance via the help of semi-supervised learning method. Experiments on house 1 and house 3 dataset of Reference Energy Disaggregation Dataset (REDD) verify the effectiveness of application of Semi-supervised learning techniques in NILM.

Abstract:Non-intrusive load monitoring (NILM) is a novel and cost-effective technology for monitoring load electricity energy consumption detail. It can support the construction of “energy internet” and electricity consumption big data in smart cities, promote the construction of internet ecology, and support the dual carbon goal achieved. Recently, most current researchers have employed machine learning methods to make those inferences. As the most challenging problem in this specific field, the machine learning algorithms usually require a large pool of labeled observations and are poor in multi-state load identification. In this paper, we first design a semi-supervised learning backbone that leverages external and internal structural information to reduce the required labeling effort. Then, a smooth teacher graph based on semi-supervised learning model is proposed for multi-state load, the teacher graph helps the fusing of cluster become tighter and more effective for multi-state load signatures. Specifically, we use the color V–I trajectory to enhance the load signature’s uniqueness. Experiments in public datasets PLAID and WHITED show the performance of the proposed method. We find that our algorithm could outperform state-of-the-art results on these datasets.

Abstract:Non-intrusive load monitoring (NILM) is a topic that lately attracts both the academic and the industrial interest. NILM is used to reveal useful information regarding the consumption breakdown on appliance or activity level, thus can be a key solution to unlock various smart-home services and opportunities. To that end, deep learning has arisen as a prominent solution. Although most of the known solutions so far focus on a predefined number of home appliances, this paper proposes a multi-class NILM system which can detect in real-time any number of appliances and can be efficiently embedded into simple microprocessors. The key feature for the identification of the appliances is the processing of measured turn-on active power transient responses sampled at 100 Hz. The NILM system includes three stages; adaptive thresholding event detection method, convolutional neural network and k-nearest neighbors classifier. For future extensions, it is capable to automatically identify new appliances; thus, no retraining and additional modeling is required.

Abstract:Energy efficiency is at a critical point now with rising energy prices and decarbonisation of the residential sector to meet the global NetZero agenda. Non-Intrusive Load Monitoring is a software-based technique to monitor individual appliances inside a building from a single aggregate meter reading and recent approaches are based on supervised deep learning. Such approaches are affected by practical constraints related to labelled data collection, particularly when a pre-trained model is deployed in an unknown target environment and needs to be adapted to the new data domain. In this case, transfer learning is usually adopted and the end-user is directly involved in the labelling process. Unlike previous literature, we propose a combined weakly supervised and active learning approach to reduce the quantity of data to be labelled and the end user effort in providing the labels. We demonstrate the efficacy of our method comparing it to a transfer learning approach based on weak supervision. Our method reduces the quantity of weakly annotated data required by up to 82.6–98.5% in four target domains while improving the appliance classification performance.

Abstract:With the proposal of the carbon peaking and neutrality targets, non-intrusive load monitoring (NILM) is crucial for energy saving and demand response. How to achieve accurate load identification (LI) is the key to the application of NILM. However, it faces a major challenge: how to identify loads accurately from massive incremental unlabeled data streams. To tackle this challenge, we propose a novel method that combines class incremental learning (CIL) and semi-supervised learning (SSL). Our method prevents catastrophic forgetting by preserving samples, distilling knowledge and aligning weights in incremental tasks. Moreover, our method leverages a semi-supervised learning structure called the Temporal Ensembling to exploit unlabeled data and overcome the semi-supervised problem in incremental learning. We test our method on PLAID and WHITED public datasets and demonstrate its effectiveness.

Abstract:Non-intrusive load monitoring (NILM) considers different approaches for disaggregating energy consumption in residential, tertiary, and industrial buildings to enable smart grid services. The main feature of NILM is that it can break down the bulk electricity demand, as recorded by conventional smart meters, into the consumption of individual appliances without the need for additional meters or sensors. Furthermore, NILM can identify when an appliance is in use and estimate its real-time consumption based on its unique consumption patterns. However, NILM is based on machine learning methods and its performance is dependent on the quality of the training data for each appliance. Therefore, a common problem with NILM systems is that they may not generalize well to new environments where the appliances are unknown, which hinders their widespread adoption and more significant contributions to emerging smart grid services. The main goal of the presented research is to apply a domain adversarial neural network (DANN) approach to improve the generalization of NILM systems. The proposed semi-supervised algorithm utilizes both labeled and unlabeled data and was tested on data from publicly available REDD and UK-DALE datasets. The results show a 3% improvement in generalization performance on highly uncorrelated data, indicating the potential for real-world applications.

Abstract:In this article, the real-time nonintrusive load-monitoring (NILM) problem with limited measurements, i.e., low sampling rate data, is investigated. NILM is a technique to identify the various types of appliances by analyzing the voltage and current features collected by sensors, such as smart outlets. It is one of the most important topics in smart grid management and optimization. Although recent NILM methods developed several general models that can be used for various scenarios, these algorithms either require high-frequency measurement devices or have been limited to use for some specific appliances. A real-time intelligent NILM algorithm that is able to be transferred among different appliances with low-frequency data is still lacking and desperately needed. In this article, a novel online learning-based intelligent NILM algorithm has been developed that can, online, infer a variety of appliances using a transferred model with limited measurements. Especially, the developed algorithm integrates the emerging transfer learning technique along with deep neural networks. Two neural networks are used in two different stages: 1) the long short-term memory (LSTM) neural network to extract the lower level spatial and temporal features from the gray-scale image generated by the measurements and 2) the probabilistic neural network (PNN) to classify the appliance type as well as transfer between appliances. Finally, the algorithm is implemented into practical smart outlet hardware to demonstrate its effectiveness.

Abstract:To achieve the goal of carbon neutrality, the demand for energy saving by the residential sector has witnessed a soaring increase. As a promising paradigm to monitor and manage residential loads, the existing studies on non-intrusive load monitoring (NILM) either lack the scalability of real-world cases or pay unaffordable attention to identification accuracy. This paper proposes a high accuracy, ultra-sparse sample, and real-time computation based NILM method for residential appliances. The method includes three steps: event detection, feature extraction and load identification. A wavelet decomposition based standard deviation multiple (WDSDM) is first proposed to empower event detection of appliances with complex starting processes. The results indicate a false detection rate of only one out of sixteen samples and a time consumption of only 0.77 s. In addition, an essential feature for NILM is introduced, namely the overshoot multiple (which facilitates an average identification improvement from 82.1% to 100% for similar appliances). Moreover, the combination of modified weighted K-nearest neighbors (KNN) and overshoot multiples achieves 100% appliance identification accuracy under a sampling frequency of 6.25 kHz with only one training sample. The proposed method sheds light on highly efficient, user friendly, scalable, and real-world implementable energy management systems in the expectable future.

Abstract:Unsafe electrical appliances pose a significant threat to life and properties. Monitoring of electrical appliances has been recognized as an important approach to improve electrical utilization safety. The purpose of this work is to detect leakage current and attribute it to an individual residential appliance in a non-intrusive way, i.e., using measurement at the electrical entry point of a home. Therefore, appliances with fault or at risk can be discovered timely without dedicated sensor installation behind the entry point. The idea is to determine whether the change of residual current is caused by a specific appliance using aggregated data. Cloud-based non-intrusive load monitoring (NILM) with load profiling is implemented to deduce detailed appliance activities and household appliance composition. Appliance leakage current can be determined by analyzing the relationship between residual current change and appliance status. The proposed approach has been verified in the lab and then deployed in a real-world residential property with all measurements integrated in the cloud. The results confirm the effectiveness of the proposed approach to detect leakage current and establish an in-depth understanding of household electrical safety.

Abstract:Intelligent power management system is an important part of the smart grid, in which the non-intrusive load monitoring technology is one of the key technologies. However, most of the load monitoring methods regard this task as a multi-classification problem, thus it is not effective to identify the unknown loads that did not participate in training. In this paper, an adaptive non-intrusive load monitoring method based on feature fusion has been proposed which utilizes both information of harmonic current feature and voltage-current (V-I) trajectory feature. The harmonic current feature is obtained from the high-frequency load sampling data through Fast Fourier Transform (FFT). At the same time, the V-I trajectory feature is obtained by using the pre-trained convolutional autoencoder neural network that was trained for feature extraction on a public dataset. After the feature extraction, the similarity between these two feature vectors and the available feature vectors in the database is calculated by TOPSIS algorithm. Then the load monitoring can be carried out according to the similarity. When the maximum similarity is greater or equal than the set threshold, the load is considered to be one of the existing loads in the database, otherwise, it will be considered as a new type of load, and the load feature database will be updated. The autoencoder model is trained by using the V-I trajectory from the BLUED dataset and the PLAID dataset is used to verify the identification accuracy of the proposed algorithm by comparison with different algorithms. On the PLAID dataset, the identification accuracy can reach above 97%. Finally, on the embedded Linux system with STM32MP1 as the core, some household electrical appliances are used for validation in real house environment. The results show that the proposed method has improved the capability of load identification by using the complementarity of different features. It can be carried out in real time on embedded system and is able to identify the unknown load at the same time.

Abstract:Nonintrusive load monitoring (NILM) involves deploying monitoring devices at the customer's bus entrance to decompose the total power captured into individual operational data for each device. Existing NILM load identification algorithms primarily adopt closed-set identification, where the same types of devices are used for both training and testing. However, a more realistic scenario is open-set identification, where device types in the training and test sets differ, encompassing not only devices from the training set but also unknown devices. To address this challenge, we propose a method leveraging reconstruction and supervised contrastive learning based on voltage–current ( – ) trajectories. Supervised contrastive learning improves the coherence of – trajectories within identical appliance classes, facilitating the model's precise comprehension and emulation of distinctive appliance behavioral patterns. By introducing an autoencoder (AE) into the model, associating each appliance class with its unique subset of features. Known – trajectories activate associated features, preserving the topological characteristics of the trajectory. In contrast, unknown – trajectories lack reconstruction mappings, resulting in thoroughly mutated trajectories. Moreover, we innovate data augmentation for contrastive learning by introducing a denoising AE (DAE). This approach introduces noise in – trajectories, the model learns to remove noise while preserving real appliance characteristics, generating more robust – trajectories. Experimental results on two publicly available datasets demonstrate the method's outstanding performance.
