Abstract:Online detection and analysis of slurry composition helps to determine the process performance of the flotation process, which is important for controlling production stability, environmental protection, and resource recovery. Our laboratory has developed a slurry analyzer based on the laser-induced breakdown spectroscopy (LIBS) technique, named SIA-LIBSlurry, which can monitor the mineral grade in slurry online. However, it is challenging to realize the high-accuracy analysis of iron grade at industrial sites due to a variety of factors, such as changes in the mineral matrix and nonlinear coupling relationships. In this article, a modeling method based on Gaussian process regression (GPR) is proposed for accurate measurement of iron grade. By designing a combination of kernel functions and noise magnitudes, the GPR model can flexibly deal with nonlinear features between data, which is suitable for the LIBS spectral data of iron ore slurries. The results showed that the GPR model achieved the best results with the highest coefficient of determination and the lowest RMSE of prediction compared with conventional quantitative analysis models such as partial least squares regression (PLS), support vector regression (SVR), and ridge regression. The DotProduct + RBF combined kernel function designed in the study better handled the linear and nonlinear relationships among the data, proving that GPR is an effective modeling method. This helps to realize the fast and effective detection of iron elements in iron ore slurry by the SIA-LIBSlurry analyzer.

A Versatile Method for Quantitative Analysis of Total Iron Content in Iron Ore Using Laser-Induced Breakdown Spectroscopy

Abstract:Focus in quality assessment of iron ore is the content of total iron (TFe). Laser-induced breakdown spectroscopy (LIBS) technology possesses the merits of rapid, in situ, real-time multielement analysis for iron ore, but its application to quantitative TFe content is subject to interference of the iron matrix effect and the lack of suitable data mining tools. Here, a new method of LIBS-based variable importance back propagation artificial neural network (VI-BP-ANN) for quantitative TFe content in iron ore was first proposed. After the LIBS spectra of 80 representative iron samples were obtained, random forest (RF) was optimized by out-of-bag (OOB) error and then used to measure and rank variable importance. The variable importance thresholds and the number of neurons were optimized with five-fold cross-validation (CV) with correlation coefficient (R2) and root mean square error (RMSE). With using only 1.40% of full spectral variables to construct BP-ANN model, the resulted R2, the root mean squared error of prediction (RMSEP) and the modeling time of the final VI-BP-ANN model was 0.9450, 0.3174 wt%, and 24 s, respectively. Compared with full spectrum-based model, for example, BP-ANN, RF, support vector machine (SVM), and PLS and VI-RF model, the VI-BP-ANN model reduced overfitting and obtained the highest R2 and the lowest RMSE both for calibration and prediction. Meanwhile, the characteristics of variables selected by VI were analyzed. In addition to the elemental emission lines of Ca, Al, Na, K, Mn, Si, Mg, Ti, Zr, and Li, partial spectral baselines of 540-610 nm and 820-970 nm were also selected as characteristic variables, which indicated that VI can take into full consideration the elemental interactions and the spectral baselines. Our approach shows that LIBS combined with VI-BP-ANN is able to quantify TFe content rapidly and accurately in iron ore.

Abstract:Due to the complexity of, and low accuracy in, iron ore classification, a method of Laser-Induced Breakdown Spectroscopy (LIBS) combined with machine learning is proposed. In the research, we collected LIBS spectra of 10 iron ore samples. At the beginning, principal component analysis algorithm was employed to reduce the dimensionality of spectral data, then we applied k-nearest neighbor model, neural network model, and support vector machine model to the classification. The results showed that the accuracy of three models were 82.96%, 93.33%, and 94.07% respectively. The results also demonstrated that LIBS with machine learning model exhibits an excellent classification performance. Therefore, LIBS technique combined with machine learning can achieve a rapid, precise classification of iron ores, and can provide a completely new method for iron ores’ selection in the metallurgical industry.

Abstract:Accurate and real-time estimation of iron ore sintering quality index is essential for the stability of the production process. However, the sintering process data is generally characterized by high dimensionality, collinearity, nonlinearity, and dynamic features, which seriously hinder the modeling performance. To cope with the complex properties mentioned above, an effective fusion of recurrent neural network with the gated recurrent unit and partial least squares (GRU-PLS) is introduced for ferrous oxide (FeO) prediction of the finished sinter. The proposed GRU-PLS model takes the advantage of conventional latent variable method but incorporates the deep inner structure between each pair of latent variables that captures the nonlinear and dynamic information simultaneously. The modeling performance of the proposed model is evaluated by the actual data collected from the iron ore sintering process in a large iron and steel group in South China. The results show the lowest prediction error of the GRU-PLS model in comparison with other counterparts. More specifically, the rootmean-square error of the GRU-PLS model is decreased by 35.29% in comparison with that for the recurrent neural network with the gated recurrent unit.

Abstract:Coal analysis is of great importance to improve coal combustion/utilization efficiency and operation safety and to reduce pollution. In this work, we develop a LIBS system for at-line coal analysis, which can pre-treat coal blocks into pressed pellets, acquire sample spectra and quantify coal properties automatically and continuously. A series of techniques are integrated in the system, including laser energy monitor and control, plasma modulation and collinear spectra collection. Moreover, the system has an integrated circuit board that is designed to precisely control the time-sequence of the hardware components; the overall design of the system ensures environmental factors are stabilised. These design considerations improve raw signal repeatability and signal-tonoise ratio. Furthermore, to improve the quantification accuracy without the use of LIBS physics knowledge, a new machine learning method is proposed, namely synergic regression (SR), which embeds a linear model in nonlinear regression. It inherits the high accuracy of nonlinear methods whilst being able to explain how specific variables contribute to the prediction. The system was demonstrated and evaluated in a real power plant for 10 weeks. The average prediction errors of calorific value (MJ/kg), sulphur (%) and volatile (%) were 0.299, 0.077 and 0.590, respectively. The evaluation demonstrated that the developed LIBS system meets the industry standards for at-line and in-situ coal analysis. Therefore, the LIBS system has significant potential impact on practices in coal utilization and similar industrial processes.

Abstract:Improving long-term stability is an important issue for large-scale applications of laser-induced breakdown spectroscopy (LIBS). Unlike laboratory instruments, many applications of LIBS instruments are in harsh outdoor environment, where instrument drift can lead to deterioration of long-term stability, hindering the application of LIBS technology to high-precision requirements. In this work, based on the designed LIBS sensor for molten steel, we analyzed the spectral drift problem of different day measurements, on the basis of which we proposed a drift correction method combining the internal standard and the dominant factor partial least squares (PLS) regression. In this method, spectra are first preprocessed to build an internal standard model of the elemental concentration ratios to spectral line intensity ratios. Then the PLS regression is utilized to construct a corrected model between the spectral intensity and the drift value of the intensity ratio. Finally, elemental concentration predictions are made by using the established internal standard model with modified spectral line intensity ratios. The method was tested on low alloy steel samples. In the experiment, the detection spectra were recorded for 9 days for quantitative analysis and drift correction of the major elements C, Si, Cr, Ni, Cu, and Mn in alloy steels. Comparing with the uncalibrated internal standard method, for the prediction of unknown samples over a long period of time, the RMSE of C, Si, Cr, Ni, Cu, and Mn were decreased by 48.74%, 50.00%, 73.30%, 72.15%, 72.57%, and 18.23%, respectively, and the RSD decreased by 27.71%, 42.97%, 35.17%, 38.95%, 55.58%, and 23.40%, respectively. Furthermore, several typical drift correction methods were also studied for comparison, and the proposed method achieved the best results on different test sets.

Abstract:The testing cycle, analyzing accuracy and precision of material ratio and chemical uniformity of sinter- ing-pelleting operation directly affect the return fines ratio and economic benefits in the steel industry. In this work, we present an in-situ measurement method, which mainly includes sample preparation, laser-induced breakdown spectroscopy (LIBS) measurement and data processing. Twelve mixture samples composed of Fe2O3, CaO and C powder materials with different concentrations were prepared and measured. The raw spectra were pre-processed with baseline, de-noise, peak finding, sum normalized, line matchning, and feature selection. Important variables of Fe, Ca and C elements were acquired and selected based on partial least squares regression coefficients (PLS-RC) and domain knowledge, and the relationship between the spectral intensity and the certified concentration information was modeled using partial least squares regression (PLSR). After data- processing, the relative standard deviation (RSD) values of Fe I (403.05 nm), Ca I (430.77 nm) and C I (247.85 nm) were optimized to be 4.20 %, 5.29 % and 7.64 %, respectively. Moreover, the coefficient of determination (R2) values of Fe, Ca and C are 98.02 %, 98.43 % and 97.18 %, respectively; the root-mean-square error (RMSE) values are 0.024, 0.010, and 0.014, respectively; and the mean absolute error (MAE) values are 0.019, 0.008, and 0.011, respectively. The evaluation demonstrated that the presented LIBS system can basically satisfy the requirement the industry standards for in-situ material ratio and uniformity analysis in sinter- ing-pelleting operation. Therefore, the proposed in-situ LIBS measuring method has great development potential and is widely applied in sintering-pelleting operations and similar processes.
Quantitative Analysis of Steel Alloy Elements Based on LIBS and Deep Learning of Multi-Perspective Features

Abstract:The Si and Mn contents in steel alloys are important characteristic indexes that influence the plasticity and welding properties of these alloys. In this work, the quantitative analysis methods for trace elements under complex alloy matrices by laser-induced breakdown spectroscopy (LIBS) are studied, which provide a foundation for utilizing LIBS technology in the rapid online detection of steel alloy properties. To improve the quantitative analysis accuracy of LIBS, deep learning algorithm methods are introduced. Given the characteristics of LIBS spectra, we explore multi-perspective feature extraction and backward differential methods to extract the spatio-temporal characteristics of LIBS spectra. The Text Convolutional Neural Network (TextCNN) model, combined with multi-perspective feature extraction, displays good stability and lower average relative errors (6.988% for Si, 6.280% for Mn) in the test set compared to the traditional quantitative analysis method and deep neural network (DNN) model. Finally, the backward differential method is employed to optimize the two-dimensional LIBS spectral input matrix, and the results indicate that the average relative errors of Si and Mn elements in the test set decrease to 5.139% and 3.939%, respectively. The method proposed in this work establishes a theoretical basis and technical support for precise prediction and online quality monitoring.

Abstract:This paper introduced electrostatic-assisted laser-induced breakdown spectroscopy (LIBS) to enhance spectral intensity and improve quantitative accuracy of trace metal elements (Cu, Al, Zn, Ca and Na) in aqueous solutions. Firstly, the effect of the voltage and pole-plate distance of electrostatic field on the spectral intensity was investigated. The spectral intensity of metal elements was enhanced by changing DC voltage and plate distance. Secondly, the effect of electrostatic-assisted LIBS on the quantitative analysis was investigated, and the limits of detection (LOD) and quantification (LOQ) were calculated with and without electrostatic-assisted LIBS. The use of electrostatic-assisted LIBS reduced the LOD and LOQ of metal elements by an order of magnitude, respectively. Finally, several regression analysis models including least squares regression analysis (PLSR), support vector machine regression analysis (SVR), backpropagation neural network regression analysis (BP-ANN), whale optimization algorithm-SVR (WOA-SVR), and whale optimization algorithm-BP (WOA-BP) were established to predict the concentration regression based on the collected spectral information. Compared to the traditional regression methods, the improved machine-learning algorithms based on intelligent optimization algorithms achieved the highest regression prediction accuracy of 99.81%. These findings confirm the capability and accuracy of electrostatic-assisted LIBS combined with machine-learning algorithms for detecting trace metal elements in aqueous solutions.

Abstract:The existence of the background signal is one of the factors leading to the uncertainty of spectral intensity, which dramatically affects the stability, repeatability, and quantitative accuracy of laser-induced breakdown spectroscopy (LIBS) measurements. In this work, the polarization-resolved LIBS (PR-LIBS) and partial least squares (PLS) regression models were proposed to improve the stability and accuracy of qualitative and quantitative analysis of steel alloy elements. The obtained spectra were pre-processed to select an appropriate number of variables, and the relationship between the spectral intensity and the certified concentration information of steel alloy samples was modeled using PLS. Compared to LIBS measurements, the relative standard deviation (RSD) and root-mean-square error (RMSE) of PR-LIBS decreased, while the signal-to-background ratio (SBR) and coefficient of determination (R2) increased. Finally, the quantitative results of LIBS and PR-LIBS of Si, Mn, Cr, and Ni in steel alloy samples using PLS were displayed and discussed. For the PR-LIBS dataset, the R2 has increased by at least 3.4%, and the root mean square error of calibration (RMSEC) and root mean square error of prediction (RMSEP) have improved by at least 6.3% and 19.0%, respectively. These findings coupled with the simplicity of the experimental process indicate that PR-LIBS is a simple and low-cost solution that can increase the stability and accuracy of LIBS measurements.

Abstract:Laser-induced breakdown spectroscopy (LIBS) technique is widely used to analyze the composition and the concentration of elements in materials,which is based on the atomic excitation and emission spectrum.It has many advantages,such as rapid,multi-element simultaneous detection and without sample pretreatment.In this paper,research progress on the application of metal element detection in such fields as alloy,soil,water,and food is reviewed.It is considered that there are some problems in this technology at present,such as low detection accuracy,poor repeatability,unstable detection signal.It is also found that the research and development of LIBS based metal element detection instrument should be developed towards the direction of conventional,portable and high precision.

Study on the Data Processing Method Applied to Improve Spectral Stability of Laser Induced Breakdown Spectroscopy in Soil Analysis

Abstract:This paper studied the data process methods of Laser-Induced Breakdown Spectroscopy (LIBS) and proposed a spectral intensity correction method utilizing laser energy monitoring and plasma morphology imaging, combined with neural network algorithm to improve the spectral stability. We set up a LIBS system, which had a laser beam sampling module to monitor laser output energy and a CMOS camera imaging module to capture plasma flame outlines. A back propagation neural network (BPNN) model was designed for standardizing the spectrum to a lower relative standard deviation (RSD) of emission line intensities, in which training spectrum, sample energy and image parameters were inputs, and the average of all the training spectrums were outputs. This method was applied in both aluminum and soil LIBS tests, and got effective results in reducing spectral intensity fluctuations. This data processing method not only provided a practical access to acquire stable spectrum information for both qualitative and quantitative LIBS analysis but also showed a bright future of combining LIBS data processing with machine learning methods.
Accurate Quantitative Analysis of LIBS With Image Form Spectra by Using a Hybrid Deep Learning Model of a Convolutional Block Attention Module-Convolutional Neural Network-Long Short-Term Memory

Abstract:With the development of miniaturized laser-induced breakdown spectroscopy (LIBS) instruments, the desire for accuracy and stability of quantitative analysis of portable LIBS systems is growing. In this research, a hybrid deep learning model of a convolutional block attention module combined with a convolutional neural network and a long short-term memory (CBAM-CNN-LSTM) was for the first time used for quantitative analysis in a LIBS system with a portable spectrometer. Among them, the spectra collected by LIBS were in the form of the image, the convolutional neural network (CNN) module was responsible for feature extraction of image spectra and mining deep features through the CBAM, and the simultaneous accurate quantitative analysis of Ca, Mg, Na, and Ba was realized by the long short-term memory (LSTM) module. Meanwhile, a linear regression (LR), a CNN, and a CNN-LSTM model were compared to the CBAM-CNN-LSTM model. The results showed that the performance of this model was much better than the LR model. More importantly, compared to CNN and CNN-LSTM, the average relative error (RE) of CBAM-CNN-LSTM was reduced by 80.5% and 68.1%, the average root mean square error (RMSE) was reduced by 56.7% and 53.4%, and the average stability was increased by 62.3% and 58.8%, respectively. In addition, the feature visualization results of CNN-LSTM and CBAM-CNN-LSTM displayed that CBAM can more effectively extract the features of characteristic peaks of corresponding elements and suppress the irrelative features. It indicated that the model can achieve an accurate and stable quantitative analysis of LIBS, which has the potential to be applied in the in- site analysis.

Abstract:Laser induced breakdown spectroscopy is an emerging elemental analytical technique with the advantage of fast response, minimal sample preparation and multi-element analysis capacities. This work studied practical use of LIBS for rapid quantification of 4 (Cu, Ni, Cr, Pb) heavy metal elements in 169 agricultural soil samples. The objective is to conclude an appropriate method to reduce the interference of matrix effect in soils within the scope of data analysis, by comparing several univariate and multivariate methods of LIBS data interpretation (full spectrum and emission lines). The proposed multivariate methods, such as the least absolute shrinkage and selection operator and principal components regression were found to be effective in reducing the matrix interference and the predictive performance was stable in our experiment, approaching normalized root mean squared error of 6.84%, 8.87%, 9,71%, 10.76% for Cu, Ni, Cr and Pb, respectively. Meanwhile, the performance of univariate analysis suffered from such effect. The results showed the importance of utilizing proper multivariate chemometrics for LIBS data interpretation when quantifying the heavy metals in soils.
Enhancement of spectral model transferability in LIBS systems through LIBS-LIPAS fusion technique

Abstract:Background: Laser-induced breakdown spectroscopy (LIBS) is extensively utilized a range of scientific and industrial detection applications owing to its capability for rapid, in-situ detection. However, conventional LIBS models are often tailored to specific LIBS systems, hindering their transferability between LIBS subsystems. Transfer algorithms can adapt spectral models to subsystems, but require access to the datasets of each subsystem beforehand, followed by making individual adjustments for the dataset of each subsystem. It is clear that a method to enhance the inherent transferability of spectral original models is urgently needed. Results: We proposed an innovative fusion methodology, named laser-induced breakdown spectroscopy fusion laser-induced plasma acoustic spectroscopy (LIBS-LIPAS), to enhance the transferability of support vector machine (SVM) original models across LIBS systems with varying laser beams. The methodology was demonstrated using nickel-based high-temperature alloy samples. Here, the area-full width at half maximum (AFCEI) Composite Evaluation Index was proposed for extracting critical features from LIBS. Further enhancing the transferability of the model, the laser-induced plasma acoustic signal was transformed from the time domain to the frequency domain. Subsequently, the feature-level fusion method was employed to improve the classification accuracy of the transferred LIBS system to 97.8 %. A decision-level fusion approach (amalgamating LIBS, LIPAS, and feature-level fusion models) achieved an exemplary accuracy of 99 %. Finally, the adaptability of the method was demonstrated using titanium alloy samples. Significance and novelty: In this work, based on plasma radiation models, we simultaneously captured LIBS and LIPAS, and proposed the fusion of these two distinct yet origin-consistent signals, significantly enhancing the transferability of the LIBS original model. The methodology proposed holds significant potential to advance LIBS technology and broaden its applicability in analytical chemistry research and industrial applications.

Abstract:Studying efficient and accurate soil heavy-metal detection technology is of great significance to establishing a modern system for monitoring soil pollution, early warning and risk assessment, which contributes to the continuous improvement of soil quality and the assurance of food safety. Laser-induced breakdown spectroscopy (LIBS) is considered to be an emerging and effective tool for heavy-metal detection, compared with traditional detection technologies. Limited by the soil matrix effect, the LIBS signal of target elements for soil heavy-metal detection is prone to interference, thereby compromising the accuracy of quantitative detection. Thus, a series of signal-enhancement methods are investigated. This study aims to explore the effect of conductive materials of NaCl and graphite on the quantitative detection of lead (Pb) in soil using LIBS, seeking to find a reliable signal-enhancement method of LIBS for the determination of soil heavy-metal elements. The impact of the addition amount of NaCl and graphite on spectral intensity and parameters, including the signal-to-background ratio (SBR), signal-to-noise ratio (SNR), and relative standard deviation (RSD), were investigated, and the mechanism of signal enhancement by NaCl and graphite based on the analysis of the three-dimensional profile data of ablation craters and plasma parameters (plasmatemperature and electron density) were explored. Univariate and multivariate quantitative analysis models including partial least-squares regression (PLSR), least-squares support vector machine (LS-SVM), and extreme learning machine (ELM) were developed for the quantitative detection of Pb in soil with the optimal amount of NaCl and graphite, and the performance of the models was further compared. The PLSR model with the optimal amount of graphite obtained the best prediction performance, with an Rp that reached 0.994. In addition, among the three spectral lines of Pb, the univariate model of Pb I 405.78 nm showed the best prediction performance, with an Rp of 0.984 and the lowest LOD of 26.142 mg/kg. The overall results indicated that the LIBS signal-enhancement method based on conductive materials combined with appropriate chemometric methods could be a potential tool for the accurate quantitative detection of Pb in soil and could provide a reference for environmental monitoring.

Abstract:It is still challenging to apply laser-induced breakdown spectroscopy (LIBS) to slurry on-stream analysis due to the moisture in slurry samples causing the low spectral intensity. In this work, a high-frequency pulsed fiber laser was proposed to quickly remove the moisture in slurry samples at the detection point for the first time. The spectral emission intensity and line broadening due Stark effect were investigated for the dual-pulse of fiber laser assisted LIBS (FL-LIBS) mode and signal-pulse LIBS (SP-LIBS) mode. It found that the spectral intensities of Fe and Ca elements were enhanced, while the matrix elements of H and O elements were decreased. Moreover, the currently available spectroscopic diagnostics of plasma, such Boltzmann plot have been used to measure the plasma temperature, while the hydrogen line broadening have been used in the characterization of electron densities. It reveals the type of higher-temperature and lower-density plasma was obtained. The experimental results demonstrated that the fiber laser had the potential to improve LIBS signal intensity and spectral resolution for aqueous matrix samples.

Abstract:Laser-induced breakdown spectroscopy(LIBS)is an emerging atomic spectroscopy technique that has the advantages of low sample pre-treatment and rapid,in situ,and simultaneous multi-element measurements.LIBS demonstrates good prospects in the field of coal analysis.In recent years,chemometric and machine learning models have been widely used to improve the quantitative accuracy of LIBS in coal analysis.Generally,these models rely on a certain number of training samples to ensure the reliability of the prediction results.However,obtaining the certified content(label information)of coal samples used for model training requires traditional chemical analysis,which is complex and time-consuming.This may lead to insufficient training samples and poor model performance.To tackle the small sample problem in LIBS-based coal analysis,this work proposes a semi-supervised learning method based on the ensemble of multiple models.5 baseline models are first established based on the initial training set,including multiple linear regression(MLR),partial least squares regression(PLSR),locally weighted partial least squares regression(LW-PLSR),support vector regression(SVR),and kernel extreme learning machine(K-ELM).The unlabelled data are processed using the 5 models,and 5 prediction values are obtained.For each unlabelled sample,the standard deviation of the 5 prediction values is calculated,and the unlabelled sample corresponding to the smallest standard deviation is added to the training set.Its pseudo label is the average of the 5 prediction values.As the training set is iteratively expanded,its corresponding training model is updated.The final training model is optimized and used to analyse the test samples.The proposed method is tested on a coal dataset containing 20 training samples,39 test samples and 280 unlabelled samples.The results show that the proposed method improves the coefficient of determination(R2)for content prediction of fixed carbon,ash,and volatile by 0.033,0.102 and 0.118,respectively.Therefore,if the number of training samples is insufficient,semi-supervised learning can effectively improve the accuracy and reliability of LIBS quantification.

Abstract:Deep learning method is applied to spectral detection due to the advantage of not needing feature engineering. In this work, the deep neural network (DNN) model is designed to perform data mining on the laser-induced breakdown spectroscopy (LIBS) spectra of the ore. The potential of heat diffusion for an affinity-based transition embedding model is first used to perform nonlinear mapping of fully connected layer data in the DNN model. Compared with traditional methods, the DNN model has the highest recognition accuracy rate (75.92%). A training set update method based on DNN output is proposed, and the final model has a recognition accuracy of 85.54%. The method of training set update proposed in this work can not only obtain the sample labels quickly but also improve the accuracy of deep learning models. The results demonstrate that LIBS combined with the DNN model is a valuable tool for ore classification at a high accuracy rate.
