Time series forecasting of pedestrian-level urban air temperature by LSTM: Guidance for practitioners

Abstract:Forecasting urban air temperature (Ta) is crucial due to its substantial socio-economic and environmental implications. Machine learning approaches, particularly neural networks with long short-term memory (LSTM), have become popular for modelling sequential data and are increasingly applied in time series tasks such as Ta forecasting. However, in practical applications, the strategies for input data and the appropriate manners for hyperparameter tuning still remain largely unclear, posing great challenges for practitioners. This study involves an extensive hyperparameter search with 21,600 trails and evaluates the spatiotemporal performance of LSTMs in forecasting Ta at pedestrian level up to 120-hour ahead, based on data from six urban weather stations in Hong Kong. Two broad categories of data input strategies were assessed, including adding auxiliary timestamp predictors and integrating external decomposition models. Both strategies significantly enhance performance, achieving over 5% reduction in root mean squared error (RMSE) compared to only using Ta series. Further analysis of hyperparameters elucidates the entire optimization landscape of LSTM, highlighting that a simple architecture with one-layer and uni-direction yields optimal performance. The findings from this study offer detailed guidance on configuring LSTMs and deepen our understanding of both the capacities and limitations of data-driven Ta forecasting.
