Abstract:Objective: Pine nuts are of great nutritional and medicinal value, but they cannot avoid such defects as mildew and insect-eating during storage. Because of their hard shells, the internal quality detection of pine nuts is a major problem for industrial sorting. For this reason, it is of great significance to carry out rapid nondestructive detection of the internal quality of pine nuts.Methods: In this paper, a rapid and nondestructive detection of pine nuts for mildew and plumpness based on terahertz transmission imaging technology was carried out. Firstly, the terahertz transmission images of pine nut samples were acquired and the terahertz spectral signals of four different regions of interest were extracted for analysis. Secondly, in order to reduce the interference of external environment on the acquisition of terahertz spectra, the terahertz spectra were pre-processedby several methods, such as ALS, AirPLS, BEADS and SNV + Detrending, and then three qualitative discriminant models, namely, Linear Discriminant Analysis (LDA), Support Vector Machine (SVM) and XGBoost integration learning, were established respectively to explore the optimal qualitative discriminant model for the detection of pine nut quality. Finally, the terahertz transmission image of pine nuts was subjected to image processing. The main feature gamut extraction combined with channel separation strategy were adopted. and then the automatic threshold segmentation algorithm was applied to perform binary threshold segmentation on the separated image, thus the plumpness of the pine nuts was calculated by calculating the ratio of the pixel points of the shell and the kernel.Results: The prediction set of BEADS + XGBoost model was established after data preprocessing with the optimal effect and the accuracy of 98.61%. The acquired terahertz images of pine nuts were extracted by the main feature gamut and the images of channel B were extracted by using channel separation. Finally, the automatic threshold segmentation of channel B was performed by using the maximum one-dimensional entropy, which can well realize the visual detection of the inner shell kernel of pine nuts.Conclusion: Terahertz imaging technology can achieve rapid and nondestructive detection of pine mildew as well as pine nut plumpness. This study provides a new rapid and nondestructive effective method for pine nut quality detection, which can provide technical reference for other shelled nut quality detection and has significant practical value.
Quality Tracing of Peanuts Using an Array of Metal-Oxide Based Gas Sensors Combined with Chemometrics Methods

Abstract:Quality tracing models were set up for both unshelled peanuts and peanut kernels by applying an array of 18 metal-oxide (MOX) based gas sensors. Acid value, peroxide value and content of crude fat of the peanuts at different storage times were measured by traditional methods as a reference. Classification results for both unshelled peanuts and peanut kernels at different storage times based on Linear Discriminant Analysis (LDA) and Support Vector Machine (SVM) were acceptable Storage time, acid value, peroxide value and content of crude fat of peanuts were predicted by Partial Least Squares Regression (PLSR) and SVM on the basis of different normalized datasets. Original datasets, datasets normalized in [0,1] and in [1,1] were considered. PLSR and SVM provided better prediction results when normalized in [0,1] and [-1,1], respectively. Correlations between adulterated levels (stale peanuts blended in fresh peanuts at levels of 0%, 25%, 50%, 75% and 100%) and sensor signals were researched by PLSR and SVM. It was found that the sensor signals and adulterated levels exhibited good correlation (R-2 > 0.801 for training and testing sets by both methods). Meanwhile, The R-2 for training and testing sets were 0.941 and 0.896 by applying SVM, respectively, and both of them were correspondingly higher than the R-2 for training and testing sets by PLSR (training: R-2=0.812; testing: R-2=0.802). The research indicates that the 18 MOX based gas sensors combined with appropriate chemometrics methods can be used as a non-destructive method in detecting peanut quality. (C) 2017 Elsevier B.V. Abstract:In this study, the changes in the quality of unshelled peanuts and peanut kernels during storage were analyzed using an electronic nose (e-nose). The physicochemical indexes (acid and peroxide values) of peanut kernels were tested by traditional method as a reference. The storage time of peanut kernels increases from left to right in the cluster analysis plot based on the physicochemical indexes. The "maximum values", "area values", and "70th s values" methods were applied to extract the feature data from the e-nose responses. Principal component analysis (PCA) results indicated that the "70th s values" method produced the most accurate results, furthermore, unshelled peanut and peanut kernel samples presented similar characteristics in the PCA plots; the partial least squares regression (PLSR) results showed that the features of unshelled peanuts and peanut kernels are highly correlated with acid and peroxide values, respectively.
A Portable NIR-system for Mixture Powdery Food Analysis Using Deep Learning

Abstract:The combination of near-infrared spectroscopy and machine intelligence has been an emerging nondestructive tool for powdery food evaluation. In this research, a novel portable system (defined as NIR-Spoon) was presented for simultaneously evaluating the mixing proportion of multi-mixture powdery food. Convolutional neural networks for multi-regression (CNN-MR) and that for feature selection (CNN-FS) were proposed for spectra processing. Multi-mixture powder samples, which contained one or more components including milk, rice, corn and wheat, were inspected by the NIR-Spoon. Results showed that the partial least squares regression (PLSR) model estimated the proportion of mixture with root mean square error (RMSE) of 0.059 and correlation coefficient (R2) of 0.938. The proposed CNN-MR realized a further improvement comparing to the benchmark PLSR method, with 0.035 for RMSE and 0.976 for R2. The CNN-MR still kept R2 of 0.970 based on 25 features selected by the CNN-FS algorithm. Moreover, the integrated load sensor could convert the proportion to the weight of each component. All hardware and software were integrated on the NIR-Spoon. Overall, the NIR-Spoon provided satisfactory accuracy and user-friendly mobile applications. It also has excellent potential to be extended for inspecting other kinds of food products in future research.

Abstract:In this research, an embedded metal oxide semiconductor (MOS) electronic nose (e-nose) was designed to detect Chinese pecan quality. To improve the performance of e-nose, three types of features were extracted to form initial feature matrix, including mean-differential coefficient value, stable value, and response area value. Furthermore, followed by the non-search feature selection strategy, optimized feature matrix was obtained through the procedure of mean analysis, variation coefficient analysis, cluster analysis and correlation analysis. It was observed that pecans were better classified after the optimization of initial feature matrix, shown by principal component analysis (PCA) score plot. And also the regression models of optimized feature matrix established by partial least squares regression (PLSR) (R-2 = 0.9377) and back propagation neural networks (BPNN) (R-2 = 0.9787) presented a better prediction capacity than these of initial one (PLSR: R-2 = 0.8887; BPNN: R-2 = 0.9093). Abstract:Rapid identification of peanut seed quality is crucial for public health. In this study, we present a terahertz wave imaging system using a convolutional neural network (CNN) machine learning approach. Terahertz waves are capable of penetrating the seed shell to identify the quality of peanuts without causing any damage to the seeds. The specificity of seed quality on terahertz wave images is investigated, and the image characteristics of five different qualities are summarized. Terahertz wave images are digitized and used for training and testing of convolutional neural networks, resulting in a high model accuracy of 98.7% in quality identification. The trained THz-CNNs system can accurately identify standard, mildewed, defective, dried and germinated seeds, with an average detection time of 2.2 s. This process does not require any sample preparation steps such as concentration or culture. Our method swiftly and accurately assesses shelled seed quality non-destructively.

Abstract:In this study, a novel uniform manifold approximation and projection combined-improved simultaneous optimization genetic algorithm-convolutional neural network (UMAP-ISOGA-CNN) algorithm was proposed. The improved simultaneous optimization genetic algorithm (ISOGA) combined with convolutional neural network (CNN) to optimize the architecture, hyperparameters, and optimizer of the CNN model simultaneously. Additionally, a uniform manifold approximation and projection (UMAP) method was used to visualize the feature space of all feature layers of the ISOGA-CNN model. The UMAP-ISOGA-CNN algorithm combined with visible and near-infrared hyperspectral imaging was used to identify peanut kernels contaminated with Aspergillus flavus and to distinguish their storage time, which is essential for the food industry to monitor the freshness of products. Overall, the UMAP-ISOGA-CNN algorithm provides useful insights into the feature space of the ISOGA-CNN model, contributing to a better understanding of the model's internal mechanisms. This study has practical implications for the food industry and future research on deep learning optimization.

Abstract:The global demand for protein is on an upward trajectory, and peanut protein powder has emerged as a significant player, owing to its affordability and high quality, with great future market potential. However, the industry currently lacks efficient methods for rapid quality testing. This research paper addressed this gap by introducing a portable device with employed near-infrared spectroscopy (NIR) to quickly assess the quality of peanut protein powder. The principal component analysis (PCA), partial least squares (PLS), and generalized regression neural network (GRNN) methods were used to construct the model to further enhance the accuracy and efficiency of the device. The results demonstrated that the newly established NIR method with PLS and GRNN analysis simultaneously predicted the fat, protein, and moisture of peanut protein powder. The GRNN model showed better predictive performance than the PLS model, the correlation coefficient in calibration (Rcal) of the fat, the protein, and the moisture of peanut protein powder were 0.995, 0.990, and 0.990, respectively, and the residual prediction deviation (RPD) were 10.82, 10.03, and 8.41, respectively. The findings unveiled that the portable NIR spectroscopic equipment combined with the GRNN method achieved rapid quantitative analysis of peanut protein powder. This advancement holds a significant application of this device for the industry, potentially revolutionizing quality testing procedures and ensuring the consistent delivery of high-quality products to fulfil consumer desires.

Abstract:Chinese pecans (Carya cathayensis) are prone to rancidity because of the high content of polyunsaturated fatty acids. It is difficult to use traditional methods to detect rancid pecan kernels without breaking the shells. In this study, an electronic nose (E-nose) was applied to detect the internal quality changes of Chinese pecans during storage. The physicochemical indexes (acid value and peroxide value) of pecan kernels were measured by traditional methods as reference. Linear discriminant analysis (LDA) was used to evaluate the classification performances of different feature extraction methods (i.e., the "10th s values", the "maximum values", the "minimum values", the "difference values", the "average values", the "area values" and the "75th s values"), and the result indicated that the "75th s values" method had the best classification performance with the first two scores explaining 97.66% of the variations. BP neural network (BPNN), learning vector quantization (LVQ), random forests (RF) and voting method were employed for further qualitative classification and the result showed that voting method performed better in classification with the 100% accuracy rate of calibration set and validation set than other three methods. Partial least squares regression (PLSR) was used for quantitative regression of acid values and peroxide values of pecan kernels, and the result provided evidences that the response data of the E-nose had a high correlation with the internal qualities of pecans. Rapid nondestructive detection of peanut varieties and peanut mildew based on hyperspectral imaging and stacked machine learning models

Abstract:Moldy peanut seeds are damaged by mold, which seriously affects the germination rate of peanut seeds. At the same time, the quality and variety purity of peanut seeds profoundly affect the final yield of peanuts and the economic benefits of farmers. In this study, hyperspectral imaging technology was used to achieve variety classification and mold detection of peanut seeds. In addition, this paper proposed to use median filtering (MF) to preprocess hyperspectral data, use four variable selection methods to obtain characteristic wavelengths, and ensemble learning models (SEL) as a stable classification model. This paper compared the model performance of SEL and extreme gradient boosting algorithm (XGBoost), light gradient boosting algorithm (LightGBM), and type boosting algorithm (CatBoost). The results showed that the MF-LightGBM-SEL model based on hyperspectral data achieves the best performance. Its prediction accuracy on the data training and data testing reach 98.63% and 98.03%, respectively, and the modeling time was only 0.37s, which proved that the potential of the model to be used in practice. The approach of SEL combined with hyperspectral imaging techniques facilitates the development of a real-time detection system. It could perform fast and non-destructive high-precision classification of peanut seed varieties and moldy peanuts, which was of great significance for improving crop yields.
Identification of fungi-contaminated peanuts using hyperspectral imaging technology and joint sparse representation model

Abstract:Peanuts with fungal contamination may contain aflatoxin, a highly carcinogenic substance. We propose the use of hyperspectral imaging to quickly and noninvasively identify fungi-contaminated peanuts. The spectral data and spatial information of hyperspectral images were exploited to improve identification accuracy. In addition, successive projection was adopted to select the bands sensitive to fungal contamination. Furthermore, the joint sparse representation based classification (JSRC), which considers neighboring pixels as belonging to the same class, was adopted, and the support vector machine (SVM) classifier was used for comparison. Experimental results show that JSRC outperforms SVM regarding robustness against random noise and considering pixels at the edge of the peanut kernel. The classification accuracy of JSRC reached 99.2% and 98.8% at pixel scale, at least 98.4% and 96.8% at kernel scale for two peanut varieties, retrieving more accurate and consistent results than SVM. Moreover, fungi-contaminated peanuts were correctly marked in both learning and test images.
A Novel Framework for Analyzing Mos E-Nose Data Based on Voting Theory: Application to Evaluate the Internal Quality of Chinese Pecans

Abstract:Metal oxide semiconductor (MOS) gas sensors have been widely used in the field of electronic nose (E-nose) for detecting the simple or complex volatile compounds. The electrical signals of MOS sensor array contain the abundant "fingerprint" information of samples. In this paper, an E-nose equipped with an array of MOS sensors was applied to detect Chinese pecans nondestructively for qualitative discrimination and quantitative prediction. Traditionally, most pattern recognition methods are based on single feature, which loses much useful information. To extract more information, a voting method, which was composed of principle component analysis (PCA) results based on 5 features (i.e., the 10th second values, the 75th second values, the area values, the maximum values and the minimum values of E-nose response curves), was proposed to classify pecan samples with different storage times. For quantitative prediction, six regression models were built on random forest (RF) algorithm to predict the contents of fatty acids in pecans. The analysis results showed that the voting method classified different pecan samples with 96% accuracy rate, and the regression models had satisfying prediction performance (R-2 > 0.97 in calibration sets and R-2 > 0.95 in validation sets). These results suggest that the voting method and RF algorithm would be promising analysis method for E-nose data. (C) 2016 Elsevier B.V. All rights reserved.
Evaluation of peach quality indices using an electronic nose by MLR, QPST and BP network

Abstract:In this paper, responses of a gas sensor array were employed to establish a quality indices model evaluating the peach quality indices. The relationship between sensor signals and the firmness, the content of sugar (CS) and acidity of “Dabai” peach were developed using multiple linear regressions with stepwise procedure, quadratic polynomial step regression (QPST) and back-propagation network. The results showed that the multiple linear regression model represented good ability in predicting of quality indices, with high correlation coefficients (R2=0.87 for penetrating force CF; R2=0.79 for content of sugar CS; R2=0.81 for pH) and relatively low average percent errors (ERR) (9.66%, 7.68% and 3.6% for CF, CS and pH, respectively). The quadratic polynomial step regression provides an accurate quality indices model, with high correlation (R2=0.92, 0.87, 0.83 for CF, CS and pH, respectively) between predicted and measured values and a relatively low error (5.47%, 3.45%, 2.57% for CF, CS and pH, respectively) for prediction. The feed-forward neural network also provides an accurate quality indices model with a high correlation (R2=0.90, 0.81, 0.87 for CF, CS and pH, respectively) between predicted and measured values and a relatively low average percent error (6.39%, 6.21%, 3.13% for CF, CS and pH, respectively) for prediction. These results prove that the electronic nose has the potential of becoming a reliable instrument to assess the peach quality indices.
An Adaptive Deep Learning Method Combined with an Electronic Nose System for Quality Identification of Soybeans Storage Period

Abstract:With the extension of storage period, the nutritional components of soybeans are lost, and the quality loss is severe, but the appearance difference is not obvious. Low-quality soybeans are often misrepresented as high-quality. In this work, an adaptive deep learning approach is proposed, integrating with an electronic nose (e-nose) system, to effectively identify the quality of soybeans with different storage periods. First, the PEN3 e-nose system is applied to obtain soybeans gas information under two different storage conditions. Secondly, a multi-spaces self-attention mechanism (MSM) is proposed to selectively important features influencing the classification performance. A lightweight gas information classification network based on this attention mechanism is designed (MSM-Net). Finally, by conducting ablation experiments and comparing with state-of-the-art gas information classification methods, MSM-Net demonstrates superior classification results. Under storage temperature of 25 °C and relative humidity of 75% RH, an accuracy of 98.50%, a precision of 98.54%, and a recall of 98.48% are achieved. Under storage temperature of 25 °C and relative humidity of 45% RH, an accuracy of 96.50%, a precision of 96.62%, and a recall of 96.85% are achieved. The findings suggest that the integration of MSM-Net and the e-nose system offers an effective detection method for monitoring the quality of soybeans.

Abstract:Measurement and Control, Ahead of Print. High-quality seeds improve the germination rate. Therefore, seed selection before sowing peanuts is crucial. Current peanut seed selection methods include color sorters and sieving machines, which are efficient but lack accuracy due to their reliance on a single indicator. Manual selection is inefficient and subject to subjective influences. Although machine vision and deep learning have performed well in crops such as corn and pepper, most existing research is based on PC or MATLAB platforms, which are not portable and are prone to interference, making them unsuitable for field applications. This study developed a lightweight model for recognizing peanut seed epidermal features. The model was based on deep learning and model quantization techniques. The transfer learning method was used to use four pre-trained models, EfficientNet_b0, EfficientNetv2-b0, MobileNet_v2_35_224, and NasNet_Mobile, as feature extraction layers, the input layer was added before the feature extraction layer, and the dropout and dense layers were added after the feature extraction layer to construct a classifier. The peanut seed selection network(PSSNet) models were constructed and named PSSNet-E, PSSNet-E2, PSSNet-M, and PSSNet-N, respectively, and trained on the Huayu 22 peanut seed dataset constructed in this study. The constructed models were compressed using model quantization technology, and four quantized models were obtained, namely PSSNet-Ef, PSSNet-E2f, PSSNet-Mf, and PSSNet-Nf. Finally, PSSNet-Mf, which had the best model evaluation, was selected as the peanut selection model for this study and deployed on a prototype for testing. Compared with the unquantized model, the size of the quantized model was reduced by two-thirds and the running speed was increased by 37%. A total of 400 Huayu 22 peanut seeds were selected as test samples, and 5 selection tests were conducted.The results showed that the average accuracy was 95.3%, which met the requirements of peanut selection at the production site.

Abstract:Food quality detection is of great importance for human health and industrial production. Currently, the common detection methods are difficult to achieve the need for fast, accurate, and non-destructive detection. In this work, an electronic nose (E-nose) detection method based on the combination of Convolutional Neural Network combined with Wavelet Scattering Network (CNN-WSN) and Improved Seahorse Optimizes Kernel Extreme Learning Machine (ISHO-KELM) is proposed for identifying the quality level of a variety of food products. In the feature extraction part, the abstract features of Convolutional Neural Network (CNN) are fused with the scattering features of Wavelet Scattering Network (WSN), and the obtained CNN-WSN fusion features can characterize the original information of the food quality effectively. In the classifier design and decision-making section, chaotic mapping is used to initialize the population in the Seahorse Optimisation Algorithm (SHO), avoiding the problem that SHO may fall into local optimal solutions. The kernel parameters and regularisation coefficients of the Kernel Extreme Learning Machine (KELM) model were then optimized by improving the locomotion, predation, and reproduction behaviors of the hippocampal populations, which solved the problem of the difficult selection of the key parameters in the model, and thus improved the accuracy and generalization of the overall model. To validate the effectiveness of the proposed food quality detection model, the E-nose system was first built and milk quality data were collected independently, and then tested on two publicly available food quality datasets as well as a self-collected milk quality dataset, respectively. The experimental results show that the food quality detection method proposed in this work has good quality assessment effect on different datasets.

Lightweight Residual Convolutional Neural Network for Soybean Classification Combined With Electronic Nose

Abstract:The quality of soybeans from different growing areas is different. It is common for low-quality soybeans to fake high-quality soybeans. This paper proposes a lightweight residual convolutional neural network (LRCNN) combined with an electronic nose (e-nose) to realize soybean quality traceability. Firstly, obtain soybean gas information from different growing areas through the e-nose. Then, according to the characteristics of e-nose detection data, the grouped heterogeneous kernel-based convolution (GHConv) is proposed, which effectively reduces the number of parameters through the combination of grouping and heterogeneous convolution. Finally, the LRCNN is proposed, which reduces the number of network parameters and avoids feature degradation, realizing the high-precision identification of soybean quality differences. In the multi-model comparison, the classification accuracy of the network is 98.37%, recall is 98.20%, and precision is 98.49%. The results show that the LRCNN combined with the e-nose can effectively identify the gas information of soybeans from different growing areas, providing a new method for soybean quality traceability.
Peanut Defect Identification Based on Multispectral Image and Deep Learning

Abstract:To achieve the non-destructive detection of peanut defects, a multi-target identification method based on the multispectral system and improved Faster RCNN is proposed in this paper. In terms of the system, the root-mean-square contrast method was employed to select the characteristic wavelengths for defects, such as mildew spots, mechanical damage, and the germ of peanuts. Then, a multispectral light source system based on a symmetric integrating sphere was designed with 2% nonuniformity illumination. In terms of Faster RCNN improvement, a texture-based attention and a feature enhancement module were designed to enhance the performance of its backbone. In the experiments, a peanut-deficient multispectral dataset with 1300 sets was collected to verify the detection performance. The results show that the evaluation metrics of all improved compared with the original network, especially in the VGG16 backbone network, where the mean average precision (mAP) reached 99.97%. In addition, the ablation experiments also verify the effectiveness of the proposed texture module and texture enhancement module in peanut defects detection. In conclusion, texture imaging enhancement and efficient extraction are effective methods to improve the network performance for multi-target peanut defect detection.

Abstract:Artificial intelligence has played a significant role in the expansion of the agriculture industry in recent times by evaluating data and making recommendations for better production. An automated method for determining significant information in seed quality analysis is the peanut maturity analysis in image processing through sensory images. The majority of the time, changes in picture intensity result in feature independence and precise maturity level determination. Therefore, agricultural precision in identifying essential features is low. To address this issue, we suggest employing a Cross-Layer Multi-Perception Neural Network (CLMPNN) for hyperspectral sensory image feature observation in order to determine the optimal assessment of peanut maturity in agriculture. The sensing unit first determines the angular cascade projection's (ACP) structural dependencies for the peanut pod structure. With the aid of color-intensive saturation, the entity projection of pod growth is found using the Slicing Fragment Segmentation (SFS) technique. This generates the various entity variations by integrating relational maturity and non-maturity findings with spectral values. Next, cross-layer multi-perception neural networks are trained with hyperspectral values optimized by LSTM to distinguish between mature and immature pods. In comparison to the other system, this one does exceptionally well in precision agriculture, with a 98.6 well recall rate, a 97.3% classification accuracy, and a 98.9% production accuracy.

Abstract:In the soybean market, it is a common phenomenon that low-quality soybeans replace high-quality soybeans. At the same time, due to the influence of the natural growth environment, the quality of soybeans produced in different origins is different. An effective method for detecting the quality of soybeans should be proposed. In this work, a deep learning method is proposed to classify the gas information of soybeans from different origins, providing an effective detection method for the quality supervision of the soybean market. Firstly, a PEN3 electronic nose (e-nose) is used to collect the gas information of soybeans from five different origins. Secondly, a multi-kernels channel attention mechanism (MKCAM) is proposed to focus on the key features of deep gas information. Thirdly, this paper proposes a residual dense block-MKCAM (RDB-MKCAM) to avoid feature degradation, improving feature expression capability. The results show that compared with other gas information classification methods, RDB-MKCAM has achieved 97.80% accuracy, 97.86% precision, 96.82% recall, and 97.33% F 1 -score, obtaining the best classification performance. In conclusion, RDB-MKCAM combined with a gas sensor array effectively realizes the classification of soybean gas information from different origins and provides an effective detection method for the quality supervision of the soybean market.
