Abstract:The total viable count (TVC) of bacteria is an important indicator of meat spoilage. Therefore the objective of the present study was to explore the potential of the hyper-spectral imaging technique in connection with the least square support vector machines (LS-SVMs) for predicting the TVC of pork. In order to simplify the TVC prediction model, stepwise discrimination method was used for the original spectrum, 1-st order and 2-nd derivative spectrum respectively to select the optimal wavelengths which can characterize the gross change trend of TVC, and some key characteristics such as the (overlap) peak and turning points of those spectrum were considered also. Then we got eight optimal wavelengths (477, 509, 540, 552, 560, 609, 720 and 772 nm) and then we used the corresponding reflective spectrum data at those optimal wavelengths to construct the TVC prediction model. The ultimate model was able to predict the TVC with R-2 = 0.9236, RMSEV = 0.3279, which indicates the feasibility of using the hyper-spectral imaging technique for the detection of total viable bacteria count in pork.
Discriminant Analysis and Quantitative Study of Antibiotics in Infant Milk Powder Based on Hyperspectral Detection

Abstract:Objective: Food quality and safety has become the focus of attention for people from all walks of life. As antibiotic residues in food will cause serious harm to human health, it is necessary to realize the rapid and non-destructive detection of antibiotic residues in food. The problem of antibiotic residues is among the most urgent problems to be tackled in the quality problems of milk powder, so it is very important to conduct accurate qualitative identification and quantitative detection of antibiotics in milk powder. Method: Based on hyperspectral technology and combined with chemometrics, this research took the three common residual antibiotics (doxycycline, chlortetracycline and oxytetracycline) in milk powder as the research objects to monitor the quality of milk powder. Firstly, Samples were prepared by grinding, drying, weighing, mixing and performing successively according to the designed concentration gradient. Then, the spectral of pure sample (infant milk powder and pure antibiotic) and samples containing three types of antibiotic residues were acquired characteristics and compared. Thirdly, to establish a qualitative discriminant model for different antibiotic residues in infant milk powder, the Partial Least Squares Discriminant Analysis (PLS-DA) and Random Forest (RF) models were established to identify antibiotic residues in milk powder. Fourthly, to establish a quantitative discriminant model for antibiotic residues in infant milk powder, to simplify the models and reduce the computational complexity, three methods, namely, Successive projection Algorithm (SPA), Uninformative Variable Elimination (UVE), and Competitive Adaptive Reweighted Sampling (CARS) were used to select the wavelengths for the optimal method. Then the Least Squares Support Vector Machine (LS-SVM) model was established to conduct quantitative detection of residual antibiotics. Result: In the qualitative analysis, PLS-DA model can roughly identify three antibiotics, with an accuracy rate of 96.2 %. RF model has better effect, with an identification accuracy reaching 100 %. In the establishment of quantitative detection model, after the spectrum wavelengths of three types of milk powder samples was selected by CARS algorithm, the CARS-LS-SVM model which was established by using only 7% of the data showed good effect. Among them, the prediction set correlation coefficient Rp and Root Mean Square Error of Prediction Set (RMSEP) of milk powder samples containing aureomycin, doxycycline and oxytetracycin residues were 0.9990 and 0.08 %, 0.9996 and 0.05 %, 0.9997 and 0.04 %, respectively. The LOD(Limit of Detection) of aureomycin, doxycycline, and oxytetracycline were 2.44 & times; 10-3, 1.51 & times; 10-3, 1.2 & times; 10-3, respectively. Conclusion: The identification of infant milk powder can be well realized by using hyperspectral technology combined with RF algorithm. The LS-SVM models were established by hyperspectral technology combined with CARS algorithm can then be used to set up better quantitative determination models of antibiotic residues in infant milk powder. This research can provide a theoretical basis for the detection of antibiotics in other types of food and can guarantee food safety to a certain extent.
Detection Of Red-Meat Adulteration By Deep Spectral-Spatial Features In Hyperspectral Images

Abstract:This paper provides a comprehensive analysis of the performance of hyperspectral imaging for detecting adulteration in red-meat products. A dataset of line-scanning images of lamb, beef, or pork muscles was collected taking into account the state of the meat (fresh, frozen, thawed, and packing and unpacking the sample with a transparent bag). For simulating the adulteration problem, meat muscles were defined as either a class of lamb or a class of beef or pork. We investigated handcrafted spectral and spatial features by using the support vector machines (SVM) model and self-extraction spectral and spatial features by using a deep convolution neural networks (CNN) model. Results showed that the CNN model achieves the best performance with a 94.4% overall classification accuracy independent of the state of the products. The CNN model provides a high and balanced F-score for all classes at all stages. The resulting CNN model is considered as being simple and fairly invariant to the condition of the meat. This paper shows that hyperspectral imaging systems can be used as powerful tools for rapid, reliable, and non-destructive detection of adulteration in red-meat products. Also, this study confirms that deep-learning approaches such as CNN networks provide robust features for classifying the hyperspectral data of meat products; this opens the door for more research in the area of practical applications (i.e., in meat processing).
Qualitative and Quantitative Detection of Minced Pork Quality by Near Infrared Reflectance Spectroscopy

Abstract:The present study is concerning qualitative and quantitative detection of minced pork quality based on FT-near infrared (FT-NIR) spectroscopy and achieving the rapid approach to detecting the minced pork quality. Firstly, FT-NIR spectroscopy combined with partial least squares (PLS) and least squares-support vector machine (LS-SVM) was used for minced pork quality prediction including discrimination of the different muscle type of pig and quantitative detection of the fat, protein and moisture content of pork. The result indicated that 100% recognition ratio for calibration and 96% recognition ratio for validation were achieved by PLSDA for 4 different muscle types of pig. These two methods for chemical composition detection both have good performances in predicting fat and moisture content, the correlation coefficient for calibration and validation was all more than 0.9, but the models for protein content prediction were of less well performances, the correlation coefficients for calibration and validation, RMSEC, RMSEP and RMSECV respectively were 0.722, 0.593, 1.595, 1.550 and 1.888, respectively. The LS-SVM method is more accurate in predicting each quality index than the PLSR method. The result shows that the prediction models for fat and moisture content based on LS-SVM have a better performance with high precision, good stability and adaptability and can be used to predict the fat and moisture content of minced pork rapidly, and provide a fast approach to discrimination of the different muscle type of pig.
Potential of Deep Learning and Snapshot Hyperspectral Imaging for Classification of Species in Meat

Abstract:In the meat industry, ensuring product authenticity is important due to its impact on human diet, processing chain as well as for ensuring fair trade practices. This study aims at investigating the potential of snapshot hyperspectral imaging (HSI) and deep learning approach for red-meat classification by combining the spectral and spatial features of HSI data of red-meat products. Moreover, this study provides a comprehensive comparison between snapshot HSI and a standard line-scanning HSI system. A novel deep 3D convolution neural network (3D-CNN) model is proposed for extracting the combined features and then classifying the meat in the HSI image. An innovative graph-based post-processing method is also proposed for enhancing the prediction of the 3D-CNN approach. Results show that the 3D-CNN approach significantly enhanced the overall accuracy of state-of-the-art models. Despite limitations in the spectral information from snapshot HSI, the 3D-CNN model shows robustness in classifying red-meat with an overall accuracy of 96.9% and 97.1% for Near-Infrared (NIR) and visible (VIS) snapshot HSI, respectively. A comparison between the HSI systems revealed that state-of-the-art models are insufficient for achieving accurate classification with snapshot HSI data while the 3D-CNN achieves excellent classification accuracy on all systems by utilizing the whole image information. The current study opens the door for further research towards real-time red-meat authenticity and mobile HSI systems using snapshot HSI and deep learning models.
[Prediction of Minced Pork Quality Attributes Using Visible and Near Infrared Reflectance Spectroscopy].

Abstract:The objective of the present study was to estimate minced pork meat quality using visible and near infrared (Vis-NIR) spectroscopy. Two hundred twenty five carcasses samples from longissimus dorsi muscle were scanned over the Vis-NIR spectral range from 350 to 1 015 nm and analysed for intramuscular fat (IMF), protein and moisture according to the official methods. Wavelet transform was employed to eliminate the spectra noise. Partial least square regression (PLSR) and support vector machine (SVM) were used to develop Vis-NIR spectroscopy models for chemical composition detection. According to calibration statistics, the best model to predict intramuscular fat content was developed by SVM with the denoised spectra, the correlation coefficient was 0.889 for calibration and 0.888 for validation. For protein and moisture, the best model was achieved with the PLS method with the correlation coefficient of 0.869 and 0.881 for protein calibration and validation sets and 0.877 and 0.848 for moisture calibration and validation sets, respectively. And all the ratios of standard deviation of validation set to root mean square error of prediction (RPD) were not more than 3.0. Results indicated that it was possible to predict chemical composition in minced pork meat. As a fast predictor of meat quality using Vis-NIR spectroscopy, it is necessary to improve the precision and the robustness of the model for practice.

Abstract:Rapid discrimination of pork in Halal and non-Halal Chinese ham sausages was developed by Fourier transform infrared (FTIR) spectrometry combined with chemometrics. Transmittance spectra ranging from 400 to 4000 cm⁻¹ of 73 Halal and 78 non-Halal Chinese ham sausages were measured. Sample preparation involved finely grinding of samples and formation of KBr disks (under 10 MPa for 5 min). The influence of data preprocessing methods including smoothing, taking derivatives and standard normal variate (SNV) on partial least squares discriminant analysis (PLSDA) and least squares support vector machine (LS-SVM) was investigated. The results indicate removal of spectral background and baseline plays an important role in discrimination. Taking derivatives, SNV can improve classification accuracy and reduce the complexity of PLSDA. Possibly due to the loss of detailed high-frequency spectral information, smoothing degrades the model performance. For the best models, the sensitivity and specificity was 0.913 and 0.929 for PLSDA with SNV spectra, 0.957 and 0.929 for LS-SVM with second derivative spectra, respectively.

Abstract:This paper reports the performance of hyperspectral imaging for detecting the adulteration in red-meat species. Line-scanning images are acquired from muscles of lamb, beef, or pork. We consider the states of fresh, frozen, or thawed meat. For each case, packing and unpacking the sample with a transparent bag is considered and evaluated. Meat muscles are defined either as a class of lamb, or as a class of beef or pork. For visualization purposes, fat regions are also considered. We investigate raw spectral features, normalized spectral features, and a combination of spectral and spatial features by using texture properties. Results show that adding texture features to normalized spectral features achieves the best performance, with a 92.8% overall classification accuracy independently of the state of the products. The resulting model provides a high and balanced sensitivity for all classes at all meat stages. The resulting model yields 94% and 90% average sensitivities for detecting lamb or the other meat type, respectively. This paper shows that hyperspectral imaging analysis provides a rapid, reliable, and non-destructive method for detecting the adulteration in red-meat products.

Abstract:The evaluation of mutton adulteration faces new challenges because of mutton flavour essence, which achieves a similar flavour between the adulterant and mutton. Hence, methods for classifying and quantifying the adulterated mutton under the effect of mutton flavour essence, based on near-infrared hyperspectral imaging (NIR-HSI, 1000–2500 nm) combined with machine learning (ML) and sparrow search algorithm (SSA), were proposed in this study. After spectral preprocessing via first derivative combined with multiple scattering correction (1D + MSC), classification and quantification models were established using back propagation neural network (BP), extreme learning machine (ELM) and support vector machine/regression (SVM/SVR). SSA was further used to explore the global optimal parameters of these models. Results showed that the performance of models improves after optimisation via the SSA. SSA-SVM achieved the optimal discrimination result, with an accuracy of 99.79% in the prediction set; SSA-SVR achieved the optimal prediction result, with an RP2 of 0.9304 and an RMSEP of 0.0458 g·g−1. Hence, NIR-HSI combined with ML and SSA is feasible for classification and quantification of mutton adulteration under the effect of mutton flavour essence. This study can provide a theoretical and practical reference for the evaluation and supervision of food quality under complex conditions.

Abstract:Chicken is at risk of contaminated foodborne pathogens in the production process. Timely and nondestructive detection of foodborne pathogens in chicken is essential for food security. The study aims to explore the feasibility of developing efficient classification models for qualitative detection of Staphylococcus aureus in chicken breast using the hyperspectral imaging technique. Principal component analysis was used to process the full spectral information and three wavelength selection methods (competitive adaptive reweighted sampling, genetic algorithm, and successive projections algorithm) were applied to extract effective wavelengths. These methods were combined with the support vector machine algorithm to develop conventional classification models, respectively. In addition, a convolutional neural network model based on deep learning was designed and trained for comparison. The performance of the convolutional neural network model was significantly better than that of conventional classification models. The overall accuracy for chicken sample classifications was improved from 83.88% to 91.38%. The results demonstrated that deep learning can effectively extract spectral features and promote the application of hyperspectral imaging in foodborne pathogens detection of chicken products.
Nondestructive detection of mutton moisture content based on hyperspectral technique

Abstract:Nondestructive detection of mutton moisture content was studied by hyperspectral imaging system(1000～2500 nm).Spectral information was collected from 108 mutton samples.The original spectra were pretreated by standard normal variate,normalization,detrend correction,Savitzky-Golay,derivative and multiple scattering correction.The partial least squares regression(PLSR) model was established for original and pre-processed spectra in the whole band.The best preprocessing algorithm was the detrend correction method.The original data was pretreated by the detrend correction method,and the characteristic wavelength was selected by the correlation coefficient method.The PLSR and stepwise multiple linear regression (SMLR) model for the mutton moisture content were established.The results showed that the SMLR model had the best effect on the prediction of moisture content.The correlation coefficient(Rc)and standard error(SEC) for calibration set were 0.8597 and 0.0521 respectively,and correlation coefficient (Rp) and standard error (SEP) for predictive set were 0.8654 and 0.0387 respectively.The results showed that it is feasible to detect mutton moisture content by hyperspectral imaging technology.

Abstract:Muttons of specific geographical origin and breed are nutritious and flavorful and they have high economic value. However, substitution and adulteration are pervasive in the market. In this study, we explore hyperspectral imaging for authenticating mutton geographical origin and breed. We extracted the reflectance spectra of 400–1000 nm from the region of interest (ROI) of hyperspectral images, and we selected effective wavelengths through principal component analysis. Then, we acquired textural features from grayscale ROI images using a gray-level gradient co-occurrence matrix and screened effective variables through correlation analysis. With various features, we used support vector machines, random forest (RF), K-nearest neighbor, and convolutional neural network to develop models to identify mutton geographical origin and breed. Optimal identification was achieved using RF with the spectra of effective wavelengths and effective variables of textural features. Classification accuracies of 99.54% and 95.67% for calibration and prediction sets, respectively, were obtained. From the confusion matrix, we authenticated each mutton type with high accuracy. Hence, HSI with effective variables of multiple features coupled with RF can identify mutton geographical origin and breed accurately and provide a potential reference for a simple system that integrates multi-wavelength spectroscopy and digital imaging.

Classification of foodborne bacteria using hyperspectral microscope imaging technology coupled with convolutional neural networks‡

Abstract:Foodborne pathogens have become ongoing threats in the food industry, whereas their rapid detection and classification at an early stage are still challenging. To address early and rapid detection, hyperspectral microscope imaging (HMI) technology combined with convolutional neural networks (CNN) was proposed to classify foodborne bacterial species at the cellular level. HMI technology can simultaneously obtain both spatial and spectral information of different live bacterial cells, while two CNN frameworks, U-Net and one-dimensional CNN (1D-CNN), were employed to accelerate the data analysis process. U-Net was used for automating cellular regions of interest (ROI) segmentation, which generated accurate cell-ROI masks in a shorter timeframe than the conventional Otsu or Watershed methods. The 1D-CNN was employed for classifying the spectral profiles extracted from cell-ROI and resulted in a higher accuracy (90%) than k-nearest neighbor (81%) and support vector machine (81%). Overall, the CNN-assisted HMI technology showed potential for foodborne bacteria detection.
Deep Spectral-spatial Features of Snapshot Hyperspectral Images for Red-meat Classification

Abstract:We investigate the potential and accuracy of snapshot hyperspectral imaging for authentication and classification of red-meat species. Snapshot hyperspectral images are acquired of lamb, beef, and pork samples. We consider 13 muscles types of standard loin and leg chops. We propose a deep 3D convolution neural network (CNN) architecture for extracting and classifying spectral-spatial learned features of red-meat. We present a comparison with state-of-the-art models including partial least-square discriminant analysis and support vector machines. Our results show that the proposed 3D-CNN model outperforms the state-of-the-art models with 95.81% and 96.01% for overall accuracy and average F1score, respectively. Visualization results show that the proposed 3D-CNN model is able to convert snapshot hyperspectral image data into an intelligent representation with accurate separation between red-meat types. This study opens the door for more research towards real-time and completely portable hyperspectral imaging systems due to the ability of snapshot hyperspectral cameras to work at video rate.
Hyperspectral imaging and deep learning for quantification of Clostridium sporogenes spores in food products using 1D- convolutional neural networks and random forest model

Abstract:Clostridium sporogenes spores are used as surrogates for Clostridium botulinum, to verify thermal exposure and lethality in sterilization regimes by food industries. Conventional methods to detect spores are time-consuming and labour intensive. The objectives of this study were to evaluate the feasibility of using hyperspectral imaging (HSI) and deep learning approaches, firstly to identify dead and live forms of C. sporogenes spores and secondly, to estimate the concentration of spores on culture media plates and ready-to-eat mashed potato (food matrix). C. sporogenes spores were inoculated by either spread plating or drop plating on sheep blood agar (SBA) and tryptic soy agar (TSA) plates and by spread plating on the surface of mashed potato. Reflectance in the spectral range of 547-1701 nm from the region of interest was used for principal component analysis (PCA). PCA was successful in distinguishing dead and live spores and different levels of inoculum (102 to 106 CFU/ml) on both TSA and SBA plates, however, was not efficient on the mashed potato (food matrix). Hence, deep learning classification frameworks namely 1D- convolutional neural networks (CNN) and random forest (RF) model were used. CNN model outperformed the RF model and the accuracy for quantification of spores was improved by 4% and 8% in the presence and absence, respectively of dead spores. The screening system used in this study was a combination of HSI and deep learning modelling, which resulted in an overall accuracy of 90-94% when the dead/inactivated spores were present and absent, respectively. The only discrepancy detected was during the prediction of samples with low inoculum levels (<102 CFU/ml). In summary, it was evident that HSI in combination with a deep learning approach showed immense potential as a tool to detect and quantify spores on nutrient media as well as on specific food matrix (mashed potato). However, the presence of dead spores in any sample is postulated to affect the accuracy and would need replicates and confirmatory assays.
Fast discriminating of purity on minced mutton using electronic tongue

Abstract:Cheaper animal protein, such as Chicken as an example, has been fraudulently used as a substitute for more expensive animal proteins, like mutton and beef. The adulteration of mutton has attracted increasing attention. It requires reliable methods for the authentication of mutton adulteration. An electronic tongue with chemically modified field-effect-transistor sensors was employed to analysis the adulteration of chicken in minced mutton. The effects of sample weight on the sensor responses of electronic tongue were studied at three different extraction solutions. Analysis of variance found that the sample weight affected the responses of the sensor significantly. With the help of Principle component analysis (PCA), the optimum experimental parameters were acquired:15 g sample extracted by 100 mL KCl solution. The adulterated mutton was made by mixing mutton with chicken at levels of 0, 20%, 40%, 60%, 80%, and 100% by weight, respectively. With the optimum experimental parameters, 168 samples of adulterated mutton were detected, and the signals were analyzed by pattern recognition techniques to build models for classification of adulterated mutton with different content of chicken, and prediction of the content of chicken in minced mutton. With PCA, the adulterated mutton samples were grouped according to their content of chicken with good classification results, except that samples containing 80%and 100%chicken partially overlapped with each other. Better classification results were found when canonical discriminant analysis (CDA) was employed, as samples containing 80% and 100% chicken were clearly grouped and separated. Multiple linear regression (MLR) and Partial least square analysis (PLS) were employed to build the predictive model for the content of chicken adulterated into minced mutton. Both models could predict the adulteration with a high determination coefficient as high as 0.9925 and 0.9923, respectively. MLR was more effective for the prediction of chicken content. The E-nose proved to be a useful authentication method for meat adulteration detection for its efficiency and high accuracy.

Abstract:Identifying live foodborne bacteria is essential for ensuring food safety and preventing foodborne illnesses. This study investigated the use of hyperspectral microscope imaging and deep learning methods to accurately distinguish between live and dead foodborne bacteria based on their spectral and morphological features. Three deep learning models, Fusion-Net I, II, and III, were developed and evaluated for their ability to classify live and dead bacterial cells of six pathogenic strains, including Escherichia coli (EC), Listeria innocua (LI), Staphylococcus aureus (SA), Salmonella Enteritidis (SE), Salmonella Heidelberg (SH), and Salmonella Typhimurium (ST). The models utilized both morphological and spectral characteristics of the bacterial cells, with inputs of average spectra and 546 nm band images. Fusion-Net I achieved high accuracy in identifying live bacterial cells, with a classification accuracy of 100% for LI, SE, ST strains and over 92.9% for EC, SA, SH. Fusion-Net II and III models were even more robust, achieving 100% accuracy consistently in classifying dead cells in all six strains. Fusion-Net III also showed the ability to identify bacterial strains with 96.9% accuracy, making it a dual-task model with potential applications in identifying live foodborne bacteria prior to foodborne outbreaks. These findings suggest that the use of hyperspectral microscope imaging and deep learning methods could provide a new tool for quickly and accurately identifying bacterial viability, thereby improving the efficiency and reliability of food safety inspection.
Rapid Detection of Total Viable Count in Intact Beef Dishes Based on NIR Hyperspectral Hybrid Model

Abstract:The total viable count (TVC) of bacteria is an important index to evaluate the freshness and safety of dishes. To improve the accuracy and robustness of spectroscopic detection of total viable bacteria count in a complex system, a new method based on a near-infrared (NIR) hyperspectral hybrid model and Support Vector Machine (SVM) algorithms was developed to directly determine the total viable count in intact beef dish samples in this study. Diffuse reflectance data of intact and crushed samples were tested by NIR hyperspectral and processed using Multiplicative Scattering Correction (MSC) and Competitive Adaptive Reweighted Sampling (CARS). Kennard-Stone (KS) and Samples Set Partitioning Based on Joint X-Y Distance (SPXY) algorithms were used to select the optimal number of standard samples transferred by the model combined with root mean square error. The crushed samples were transferred into the complete samples prediction model through the Direct Standardization (DS) algorithm. The spectral hybrid model of crushed samples and full samples was established. The results showed that the Determination Coefficient of Calibration (RP2) value of the total samples prediction set increased from 0.5088 to 0.8068, and the value of the Root Mean Square Error of Prediction (RMSEP) decreased from 0.2454 to 0.1691 log10 CFU/g. After establishing the hybrid model, the RMSEP value decreased by 9.23% more than before, and the values of Relative Percent Deviation (RPD) and Reaction Error Relation (RER) increased by 12.12% and 10.09, respectively. The results of this study showed that TVC instewed beef samples can be non-destructively determined based on the DS model transfer method combined with the hybrid model strategy. This study provided a reference for solving the problem of poor accuracy and reliability of prediction models in heterogeneous samples.

Abstract:The detection of meat texture is of great value because it is the key factor that drives consumer purchasing decisions. In this study, a hyperspectral imaging (HSI) system was utilized to determine the texture parameters of Tan mutton. In order to observe the influence of mutton spectra during different refrigeration periods for modeling, hyperspectral images of the Tan mutton samples were collected in the 900–1700 nm spectral range, and the correction models of Tan mutton texture parameters were established. The four machine learning algorithms, such as partial least squares regression (PLSR), least squares support vector machine (LSSVM), random forest (RF), and decision trees (DT), were developed to establish the spectral models based on the characteristic bands selected by different extraction strategies including interval variable iterative space shrinkage approach (iVISSA), competitive adaptive reweighted sampling (CARS), successive projection algorithm (SPA) and variable combination population analysis (VCPA). The results showed that the LSSVM-iVISSA-CARS models exhibited excellent performance in predicting hardness and gumminess with root-mean-square errors (RMSEP) of 5.259 and 3.051 as well as the coefficient of determination for the prediction data set (Rp 2) of 0.986 and 0.984 respectively. Good performances were achieved with Rp 2 of 0.987 and RMSEP of 4.970 with the LSSVM-iVISSA-SPA model for chewiness, respectively. Therefore, HSI has potential for the evaluation and prediction of texture parameters in Tan mutton.

Abstract:The adulteration of pork mixed in mutton is pervasive in the market. However, when the adulterated mutton with multi-part pork is mixed, the discrimination becomes difficult due to differences in composition. Meanwhile, with the diversification of adulteration methods, food additives are also mixed into adulterated mutton to interfere with discrimination. In this study, the discrimination of mutton adulteration with multi-part pork (from back, hind leg, and front leg) under the influence of mutton flavour essence and colourant was explored using NIR-HSI. A novel framework in which three parallel convolutional neural networks (CNNs) serve as feature extractors was designed to obtain the multi-part depth fusion features of the sample. After obtaining fusion features, classification models were established by using back propagation neural network (BPNN), random forest (RF), and support vector machine (SVM). Sparrow search algorithm (SSA), genetic algorithm (GA), and particle swarm optimization (PSO) were employed for parameter optimization of classifiers. The results showed that the performance of models based on fusion features was significantly better than that of models without considering the characteristics of pork parts. The optimized SVM classifier via SSA obtained the best result. The overall accuracy, F1-score, and kappa value of the external validation set were 98.61%, 97.86%, and 96.61%, respectively. Overall, NIR-HSI combined with CNN and optimized SVM could function as a robust and accurate detection method for discriminating adulterated mutton with multi-part pork under food additives effect.
