Abstract:This research aims to improve the accuracy and efficiency of steel surface defect detection and address the current insufficient algorithm performance in steel defect detection, especially the challenges in multi-scale feature extraction and parameter efficiency. Based on the improved YOLOv8 network structure, three key improvement points are introduced: the DBB module optimizes multi-scale feature extraction, the MSCA attention mechanism enhances the model's defect detection accuracy, and the optimized GDetect module reduces the amount of parameters and calculations. Extensive experiments and comparative analysis using the NEU-DET data set verify the effectiveness of the improved method. Ablation experiments show that using DBB or MSCA alone has limited performance improvement, but when MSCA and GDetect are combined, the model has significant improvements in Precision, Recall, and mAP50 indicators. Comparative experiments show that the performance of this algorithm is close to or even surpasses some more complex models while remaining relatively lightweight. The average accuracy mean analysis for six defect categories also shows the superior performance of this algorithm for various types of defects. The steel surface defect detection method proposed in this study based on the improved YOLOv8 network has made significant progress in the field of steel defect detection. The improved method improves detection accuracy, solves common problems, and achieves high performance while maintaining lightweight, providing an efficient and feasible solution for steel surface defect detection.

Abstract:To improve the accuracy of steel surface defect detection, an improved model of multi-directional optimization based on the YOLOv8 algorithm was proposed in this study. First, we innovate the CSP Bottleneck with the two convolutions (C2F) module in YOLOv8 by introducing deformable convolution (DCN) technology to enhance the learning and expression ability of complex texture and irregular shape defect features. Secondly, the advanced Bidirectional Feature Pyramid Network (BiFPN) structure is adopted to realize the weight distribution learning of input features of different scales in the feature fusion stage, allowing for more effective integration of multi-level feature information. Next, the BiFormer attention mechanism is embedded in the backbone network, allowing the model to adaptively allocate attention based on target features, such as flexibly and efficiently skipping non-critical areas, and focusing on identifying potentially defective parts. Finally, we adjusted the loss function from Complete-Intersection over Union (CIoU) to Wise-IoUv3 (WIoUv3) and used its dynamic non-monotony focusing property to effectively solve the problem of overfitting the low quality target bounding box. The experimental results show that the mean Average Precision (mAP) of the improved model in the task of steel surface defect detection reaches 84.8%, which depicts a significant improvement of 6.9% compared with the original YOLO8 model. The improved model can quickly and accurately locate and classify all kinds of steel surface defects in practical applications and meet the needs of steel defect detection in industrial production.

Abstract:During the production process of steel, there are often some defects on the surface of the product. Therefore, detecting defects is the key to produce high-quality products. At the same time, the defects of the steel have caused huge losses to the high-tech industry. A steel surface defect detection algorithm based on improved YOLO-V7 is proposed to address the problems of low detection speed and low detection accuracy of traditional steel surface defect detection methods. First, we use the de-weighted BiFPN structure to make full use of the feature information to strengthen feature fusion, reduce the loss of feature information during the convolution process, and improve the detection accuracy. Secondly, the ECA attention mechanism is combined in the backbone part to strengthen the important feature channels. Finally, the original bounding box loss function is replaced by the SIoU loss function, where the penalty term is redefined by taking the vector angle between the required regressions into account. The experimental results show that the improved model proposed in this paper has higher performance compared with other comparison models. Based on our experiments, the proposed method yields 80.2% mAP and 81.9% on the GC10-DET dataset and NEU-DET dataset with high speed, which is better than other existing models.

Abstract:Steel, as one of the most used materials, is of great importance for steel defect detection in industry. Aiming at the existing existing deep learning-based steel surface defect detection algorithms that have problems such as misdetection, leakage, low detection accuracy and speed, a steel surface defect detection algorithm YOLOv8n-CFP is proposed to improve YOLOv8n. Firstly, the CPCA attention mechanism module is added, which combines the channel attention mechanism with the spatial attention mechanism, to improve the model's recognition accuracy and generalization ability. After that, the Faster module is used instead of Bottleneck to reduce the computational complexity of the C2f module and lighten the network structure. Finally, the PIoU loss function is used instead of CIoU to optimize the performance of anchor frame regression, which guides the anchor frame to regress efficiently and achieve faster convergence by combining the target size adaptive penalty factor and gradient adjustment function. The experiments show that compared with the basic YOLOv8n network, the YOLOv8n-CFP inspection network improves the mAP from 76.2% to 79.0% on the steel surface defects inspection dataset of YOLOv8n, which is an improvement of 2.8%, and the model volume, parameter count, and computational size are reduced by 17.5%, 18.3%, and 17.3%, respectively, and the FPS value is improved by 60.4. Compared with other YOLOv8n networks, the average accuracy mAP of YOLOv8n-CFP inspection network is increased to 79.0%. Compared with other YOLO algorithms, YOLOv8n-CFP has significant advantages in steel surface defect detection.

Abstract:The detection of surface defects on metal products during the production process is crucial for ensuring high-quality products. These defects also lead to significant losses in the high-tech industry. To address the issues of slow detection speed and low accuracy in traditional metal surface defect detection, an improved algorithm based on the YOLOv7-tiny model is proposed. Firstly, to enhance the feature extraction and fusion capabilities of the model, the depth aware convolution module (DAC) is introduced to replace all ELAN-T modules in the network. Secondly, the AWFP-Add module is added after the Concat module in the network's Head section to strengthen the network's ability to adaptively distinguish the importance of different features. Finally, in order to expedite model convergence and alleviate the problem of imbalanced positive and negative samples in the study, a new loss function called Focal-SIoU is used to replace the original model's CIoU loss function. To validate the effectiveness of the proposed model, two industrial metal surface defect datasets, GC10-DET and NEU-DET, were employed in our experiments. Experimental results demonstrate that the improved algorithm achieved detection frame rates exceeding 100 fps on both datasets. Furthermore, the enhanced model achieved an mAP of 81% on the GC10-DET dataset and 80.1% on the NEU-DET dataset. Compared to the original YOLOv7-tiny algorithm, this represents an increase in mAP of nearly 11% and 9.2%, respectively. Moreover, when compared to other novel algorithms, our improved model demonstrated enhanced detection accuracy and significantly improved detection speed. These results collectively indicate that our proposed enhanced model effectively fulfills the industry's demand for rapid and efficient detection and recognition of metal surface defects.

Abstract:Steel surface defect detection is an indispensable part of industrial production and processing processes. It helps to reduce production costs, ensure product quality, improve production safety and compliance, and maintain sustainability and competitiveness. To address the low detection accuracy of traditional methods, this paper developed and investigated an improved algorithm based on YOLO for steel surface defect detection: ECA(Efficient Channel Attention) -SimSPPF (Simplified Spatial Pooling - Fast) -SIoU (Scylla Intersection over Union) -Yolov5. First, deformable convolutions were used to replace some conventional convolutions in the model, which expanded the receptive field and improved detection accuracy. Additionally, Efficient Channel Attention was integrated into the model to improve the weight of important information. Then, the SimSPPF was employed in place of the SPP module in the model, reducing computational complexity. Finally, the SIoU loss function was utilized to handle bounding box regression more effectively. The paper conducted different ablation experiments, and the improved ECA-SimSPPF-SIoU-Yolov5 algorithm demonstrated superior detection performance. Using the NEU-DET dataset, the mAP reached 78.8%, which was a 7.1% improvement higher than the original model, while the Recall reached 76.4% and improved by 3.7% compared to the original model. The improved model showed significant improvements in terms of mAP and Recall. Furthermore, the paper conducted multiple comparative experiments, comparing the model with other attention mechanisms and loss functions. The results demonstrated that the improved ECA-SimSPPF-SIoU-Yolov5 algorithm achieved good detection results in terms of mAP and Recall. In the third comparative experiment, the model was compared with YOLOv5 model with different network depths and the latest Yolov8 model, and the improved model also achieved good detection accuracy.

Abstract:Aiming at the problems of low detection efficiency and poor detection accuracy caused by texture feature interference and dramatic changes in the scale of defect on steel surfaces, an improved YOLOv5s model is proposed. In this study, we propose a novel re-parameterized large kernel C3 module, which enables the model to obtain a larger effective receptive field and improve the ability of feature extraction under complex texture interference. Moreover, we construct a feature fusion structure with a multi-path spatial pyramid pooling module to adapt to the scale variation of steel surface defects. Finally, we propose a training strategy that applies different kernel sizes for feature maps of different scales so that the receptive field of the model can adapt to the scale changes of the feature maps to the greatest extent. The experiment on the NEU-DET dataset shows that our model improved the detection accuracy of crazing and rolled in-scale, which contain a large number of weak texture features and are densely distributed by 14.4% and 11.1%, respectively. Additionally, the detection accuracy of inclusion and scratched defects with prominent scale changes and significant shape features was improved by 10.5% and 6.6%, respectively. Meanwhile, the mean average precision value reaches 76.8%, compared with the YOLOv5s and YOLOv8s, which increased by 8.6% and 3.7%, respectively.

Abstract:To address the issue of low detection accuracy of steel surface defects due to complex texture background interference and complex defect morphology, this paper proposes an improved YOLOv8 model based on MobileViTv2 and Cross-Local Connection for steel surface defect detection. Firstly, the lightweight MobileViTv2 network is introduced into the backbone network, which enhances the feature extraction capability of the model in complex defect shapes by combining the advantages of CNN and Transformer. Then, the designed CLC method is introduced into the neck network, which connects deep and shallow features through additional convolutional layers, further integrating defect features in the presence of complex texture background interference. Finally, the NET-DET dataset is augmented to improve the model's robustness. Experimental results show that the mAP of the improved model is 74.1%, with a detection speed of 86.2 FPS and model memory usage of 27.5 MB. Compared to YOLOv5 and YOLOv8, the mAP of the improved model is increased by 6.5% and 4%, respectively. Compared to existing object detection models, the improved model has the characteristics of high detection accuracy and fast detection speed, meeting the requirements of industrial production for steel surface defect detection.

Abstract:The fast and accurate detection of steel surface defects has become an important goal of research in various fields. As one of the most important and effective methods of detecting steel surface defects, the successive generations of YOLO algorithms have been widely used in these areas; however, for the detection of tiny targets, it still encounters difficulties. To solve this problem, the first modified PP-YOLOE algorithm for small targets is proposed. By introducing Coordinate Attention into the Backbone structure, we encode channel relationships and long-range dependencies using accurate positional information. This improves the performance and overall accuracy of small target detection while maintaining the model parameters. Additionally, simplifying the traditional PAN+FPN components into an optimized FPN feature pyramid structure allows the model to skip computationally expensive but less relevant processes for the steel surface defect dataset, effectively reducing the computational complexity of the model. The experimental results show that the overall average accuracy (mAP) of the improved PP-YOLOE algorithm is increased by 4.1%, the detection speed is increased by 2.06 FPS, and the accuracy of smaller targets (with a pixel area less than 322) that are more difficult to detect is significantly improved by 13.3% on average, as compared to the original algorithm. The detection performance is also higher than that of the mainstream target detection algorithms, such as SSD, YOLOv3, YOLOv4, and YOLOv5, and has a high application value in industrial detection.

Abstract:To solve the problem of low detection accuracy caused by background interference and diverse target forms, a series of improvements are proposed to improve the detection accuracy. According to the various characteristics of steel surface defects, this paper presents the K-Means clustering algorithm to optimize the clustering results and quickly and accurately obtain the size of the prior box. In view of the small proportion of the target defect area in the overall image and background interference, a two-way attention module (TWA-Block) is proposed to establish the long-distance dependence of the spatial domain and channel domain features, and a background suppression function is designed to realize the division of defect areas. Experiments of the proposed improvements in the NEU-DET dataset based on the YOLO series model show that the detection accuracy of all the improved YOLO series models has improved, and the number of parameters will not increase substantially

Abstract:Steel is a crucial material that is extensively utilized in various aspects of daily life and holds significant importance. However, during its production, there is a possibility of certain defects arising that could have a negative impact on the quality of the steel. Only by accurately detecting the defects on the steel surface can we avoid the harm caused by defects in steel. Because the steel surface defect detection algorithm is prone to misdetection, missed detection, and other problems, a steel surface defect detection algorithm based on improved YOLOX is proposed. First, the CSPCrossLayer module proposed in this paper is used to replace the CSPLayer structure in the backbone network to enrich the gradient information of the network and strengthen the feature extraction capability; Then, the SA (Shuffle Attention) module is added after the output of the backbone network, highlighting the general information to input high-quality features for the feature fusion network; Finally, the PSblock module is proposed to replace the CSPLayer structure in the feature fusion network, which reduces redundant computations to efficiently perform feature fusion on feature layers of different scales and improves the feature fusion capability of the model. The experiments involved testing the algorithm on two datasets: the publicly available NEU-DET dataset and a steel rail dataset collected in this paper. The algorithm can reach 77% mAP on the NEU-DET dataset, while the detection speed is 100 FPS. It reaches 88.8% mAP on the steel rail dataset, and the detection speed is 93FPS. These results demonstrate that the proposed algorithm is capable of swiftly and accurately detecting surface defects in steel materials.

Abstract:The pursuit of higher recognition accuracy and speed with smaller model sizes has been a major research topic in the detection of surface defects in steel. In this paper, we propose an improved high-speed and high-precision Efficient Fusion Coordination network (EFC-YOLO) without increasing the model's size. Since modifications to enhance feature extraction in shallow networks tend to affect the speed of model inference, in order to simultaneously ensure the accuracy and speed of detection, we add the improved Fusion-Faster module to the backbone network of YOLOv7. Partial Convolution (PConv) serves as the basic operator of the module, which strengthens the feature-extraction ability of shallow networks while maintaining speed. Additionally, we incorporate the Shortcut Coordinate Attention (SCA) mechanism to better capture the location information dependency, considering both lightweight design and accuracy. The de-weighted Bi-directional Feature Pyramid Network (BiFPN) structure used in the neck part of the network improves the original Path Aggregation Network (PANet)-like structure by adding step branches and reducing computations, achieving better feature fusion. In the experiments conducted on the NEU-DET dataset, the final model achieved an 85.9% mAP and decreased the GFLOPs by 60%, effectively balancing the model's size with the accuracy and speed of detection.

SteelGuard-yolo: Steel Surface Defect Detection Network Based on Improved YOLOv5s

Abstract:Steel is playing an increasingly important role in industry, and the detection of defects on its surface is also of great significance. The complex and diverse defects on the steel surface bring great challenges to the detection. In this paper, we propose a SteelGuard-yolo based steel surface defect detection model, whose main role is to improve the existing algorithms for detecting steel surface defects. First, we design the C2f module with weight aggregation and introduce the BiFormer attention mechanism to improve the feature extraction capability of the model. Second, we design a new up-sampling structure and introduce the Multi-Scale Dilated Attention (MSDA) module to effectively improve the feature fusion capability of the model. Finally, we introduce the Simam attention mechanism and use EIoU as a new loss function to improve the robustness and accuracy of the model.SteelGuard-yolo has a powerful multi-scale feature fusion capability and achieves an ideal balance between latency and accuracy. The algorithm proposed in this paper is tested on the NEU-DET dataset and achieves an average accuracy of 69.0%, which compares favorably with most one- and two-stage detection algorithms.
Online Detection of Surface Defects Based on Improved YOLOV3

Abstract:Aiming at the problems of low efficiency and poor accuracy in the product surface defect detection. In this paper, an online surface defects detection method based on YOLOV3 is proposed. Firstly, using lightweight network MobileNetV2 to replace the original backbone as the feature extractor to improve network speed. Then, we propose an extended feature pyramid network (EFPN) to extend the detection layer for multi-size object detection and design a novel feature fusing module (FFM) embedded in the extend layer to super-resolve features and capture more regional details. In addition, we add an IoU loss function to solve the mismatch between classification and bounding box regression. The proposed method is used to train and test on the hot rolled steel open dataset NEU-DET, which contains six typical defects of a steel surface, namely rolled-in scale, patches, crazing, pitted surface, inclusion and scratches. The experimental results show that our method achieves a satisfactory balance between performance and consumption and reaches 86.96% mAP with a speed of 80.96 FPS, which is more accurate and faster than many other algorithms and can realize real-time and high-precision inspection of product surface defects.

Abstract:The surface defects of industrial structural parts have the characteristics of a large-scale span and many small objects, so a novel YOLOv3 model, the YOLOv3-ALL algorithm, is proposed in this paper to solve the problem of precise defect detection. The K-means++ algorithm is combined with the intersection-over-union (IoU) and comparison of the prior box for clustering, which improves the clustering effect. The convolutional block attention module (CBAM) is embedded in the network, thus improving the ability of the network to obtain key information in the image. By adding fourth-scale prediction, the detection capability of a YOLOv3 network for small-object defects is greatly improved. A loss function is designed, which adds the generalized intersection-over-union (GIoU) loss combined with focal loss to solve the problems of L2 loss and class imbalance in samples. Experiments regarding contour-defect detection for stamping parts show that the mean average precision (mAP) of the YOLOV3-ALL algorithm reaches 75.05% in defect detection, which is 25.16% higher than that of the YOLOv3 algorithm. The average detection time is 39 ms/sheet. This proves that the YOLOv3-ALL algorithm has good real-time detection efficiency and high detection accuracy.

Abstract:With the development of artificial intelligence technology and the popularity of intelligent production projects, intelligent inspection systems have gradually become a hot topic in the industrial field. As a fundamental problem in the field of computer vision, how to achieve object detection in the industry while taking into account the accuracy and real-time detection is an important challenge in the development of intelligent detection systems. The detection of defects on steel surfaces is an important application of object detection in the industry. Correct and fast detection of surface defects can greatly improve productivity and product quality. To this end, this paper introduces the MSFT-YOLO model, which is improved based on the one-stage detector. The MSFT-YOLO model is proposed for the industrial scenario in which the image background interference is great, the defect category is easily confused, the defect scale changes a great deal, and the detection results of small defects are poor. By adding the TRANS module, which is designed based on Transformer, to the backbone and detection headers, the features can be combined with global information. The fusion of features at different scales by combining multi-scale feature fusion structures enhances the dynamic adjustment of the detector to objects at different scales. To further improve the performance of MSFT-YOLO, we also introduce plenty of effective strategies, such as data augmentation and multi-step training methods. The test results on the NEU-DET dataset show that MSPF-YOLO can achieve real-time detection, and the average detection accuracy of MSFT-YOLO is 75.2, improving about 7% compared to the baseline model (YOLOv5) and 18% compared to Faster R-CNN, which is advantageous and inspiring.

Steel Surface Defect Detection Method Based on Improved YOLOv9 Network

Abstract:This paper introduces a new steel defect detection model CK-NET, which uses YOLOv9c as the baseline model and adopts YOLOv9's model architecture for improvement. The proposed model addresses issues of shallow information loss and insufficient feature extraction and fusion caused by network deepening. A new feature extraction module is designed to control model parameters and enhance feature extraction. Minor improvements to Convolutional Block of Attention Module (CBAM) and the introduction of deformable convolutions in the backbone network further enhance feature extraction. A new feature fusion module, combined with a self-attention mechanism (SA), elegantly fuses features from different levels to assist downstream detection tasks. The Programmable Gradient Information (PGI) auxiliary branch is also improved to better fuse features and guide model learning with gradient information. All improved modules have been integrated into CK-NET. Experiments on the NEU-DET dataset demonstrate that CK-Net achieves a 13.2% higher mAP value than YOLOv9c, reaching a 92.1% mAP value while maintaining similar model parameters, validating the model's effectiveness.

GDM-YOLO: A Model for Steel Surface Defect Detection Based on YOLOv8s

Abstract:Steel materials are extensively used across various industries. Detecting surface defects in steel strips during production processes is crucial. Existing steel surface defect detection methods exhibit inadequate accuracy and excessive computational complexity, posing challenges for real-time industrial deployment. In this paper, a novel model is designed named GDM-YOLO, specifically tailored for steel surface defect detection tasks, built upon the YOLOv8s network. Firstly, the Space-to-Depth Ghost Convolution (SPDG) downsampling module is introduced and used in the backbone network, aimed at minimizing information loss during downsampling operations while optimizing computational efficiency. Secondly, this work introduces the C2f-Dilated-Reparam-Block (C2f-DRB) module, leveraging reparameterization and large kernel convolutions to enhance feature extraction capabilities without compromising inference costs. Lastly, the novel Multiscale Feature Enhancement Block (MFEB) module was designed, to enhance the small target detection layer by integrating multi-scale feature fusion, further improving detection accuracy. Experimental results demonstrate a 3% improvement in detection accuracy on the NEU-DET dataset compared to the baseline YOLOv8s model. Our approach achieves superior detection performance while reducing parameter requirements and computational complexity, meeting the real-time demands of steel surface defect detection in industrial production.

Abstract:Aiming at the problem of low efficiency of manual detection in the field of metal surface defect detection, a deep learning defect detection method based on improved YOLOv5 algorithm is proposed. Firstly, in the feature enhancement part, we replace the multi-head self-attention module of the standard transformer encoder with the EVC module to improve the feature extraction ability. Second, in the prediction part, adding a small target detection head can reduce the negative impact of drastic object scale changes and improve the accuracy and stability of detection. Finally, the performance of the algorithm is verified by ablation experiments and analogy experiments. The experimental results show that the improved algorithm has greatly improved mAP and FPS on the data set, and can quickly and accurately identify the types of metal surface defects, which has reference significance for practical industrial applications.
