Abstract:Hyperspectral scattering techniques were used to predict beef pH, tenderness (i.e. WBSF: Warner-Bratzler Shear Force) and color parameters. Thirty-three fresh strip loin cuts were collected from 2-day postmortem carcass. After capturing scattering images and measuring pH values, the samples were vacuum packaged and aged to seventh day, then their color parameters (L*, a*, b*) and WBSF were measured as references. The optical scattering profiles were extracted from the hyperspectral images and fitted to the Lorentzian distribution (LD) function with three parameters. LD parameters, such as the peak height, full scattering width at half maximum (FWHM) and the scattering asymptotic were calculated at individual wavelength. Stepwise regression was used to determine optimal combinations of wavelengths for each of parameters. The optimal combinations were then used to establish multi-linear regression (MLR) models to predict the beef attributes. The full cross validation method was used to examine the performance of models. The models were able to predict beef WBSF with R-CV=0.86, and with the SECV(the standard error of cross validation) of 11.7 N, 91% classification accuracy could be obtained. Two-day pH values with R-CV=0.86, SECV=0.07 and color parameters (L*, a*, b*) with R-CV of 0.92, 0.90 and 0.88, with the SECV of 0.90, 1.34 and 0.41 were obtained respectively. This research provided available technique for the development of multispectral system, which could be implemented online to determine beef steaks color and tenderness.

Abstract:The quality and flavor of tea leaves are significantly influenced by chemical composition, with the content of free amino acids serving as a key indicator for assessing the quality of Tencha. Accurately and quickly measuring free amino acids during tea processing is crucial for monitoring and optimizing production processes. However, traditional chemical analysis methods are often time-consuming and costly, limiting their application in real-time quality control. Hyperspectral imaging (HSI) has shown significant effectiveness as a component detection tool in various agricultural applications. This study employs VNIR-HSI combined with machine learning algorithms to develop a model for visualizing the total free amino acid content in Tencha samples that have undergone different processing steps on the production line. Four pretreating methods were employed to preprocess the spectra, and partial least squares regression (PLSR) and least squares support vector machine regression (LS–SVR) models were established from the perspectives of individual processes and the entire process. Combining competitive adaptive reweighted sampling (CARS) and variable iterative space shrinkage approach (VISSA) methods for characteristic band selection, specific bands were chosen to predict the amino acid content. By comparing modeling evaluation indicators for each model, the optimal model was identified: the overall model CT+CARS+PLSR, with predictive indicators Rc2 = 0.9885, Rp2 = 0.9566, RMSEC = 0.0956, RMSEP = 0.1749, RPD = 4.8021, enabling the visualization of total free amino acid content in processed Tencha leaves. Here, we establish a benchmark for machine learning-based HSI, integrating this technology into the tea processing workflow to provide a real-time decision support tool for quality control, offering a novel method for the rapid and accurate prediction of free amino acids during tea processing. This achievement not only provides a scientific basis for the tea processing sector but also opens new avenues for the application of hyperspectral imaging technology in food science.
On-line prediction of fresh pork quality using visible/near-infrared reflectance spectroscopy.

Abstract:Visible/near-infrared (Vis/NIR) spectroscopy was tested to predict the quality attributes of fresh pork (content of intramuscular fat, protein and water, pH and shear force value) on-line. Vis/NIR spectra (350–1100nm) were obtained from 211 samples using a prototype. Partial least-squares regression (PLSR) models were developed by external validation with wavelet de-noising and several pre-processing methods. The 6th order Daubechies wavelet with 6 decomposition levels (db6–6) showed high de-noising ability with good information preservation. The first derivative of db6–6 de-noised spectra combined with multiplicative scatter correction yielded the prediction models with the highest coefficient of determination (R2) for all traits in both calibration and validation periods, which were all above 0.757 except for the prediction of shear force value. The results indicate that Vis/NIR spectroscopy is a promising technique to roughly predict the quality attributes of intact fresh pork on-line.
[Prediction of Minced Pork Quality Attributes Using Visible and Near Infrared Reflectance Spectroscopy].

Abstract:The objective of the present study was to estimate minced pork meat quality using visible and near infrared (Vis-NIR) spectroscopy. Two hundred twenty five carcasses samples from longissimus dorsi muscle were scanned over the Vis-NIR spectral range from 350 to 1 015 nm and analysed for intramuscular fat (IMF), protein and moisture according to the official methods. Wavelet transform was employed to eliminate the spectra noise. Partial least square regression (PLSR) and support vector machine (SVM) were used to develop Vis-NIR spectroscopy models for chemical composition detection. According to calibration statistics, the best model to predict intramuscular fat content was developed by SVM with the denoised spectra, the correlation coefficient was 0.889 for calibration and 0.888 for validation. For protein and moisture, the best model was achieved with the PLS method with the correlation coefficient of 0.869 and 0.881 for protein calibration and validation sets and 0.877 and 0.848 for moisture calibration and validation sets, respectively. And all the ratios of standard deviation of validation set to root mean square error of prediction (RPD) were not more than 3.0. Results indicated that it was possible to predict chemical composition in minced pork meat. As a fast predictor of meat quality using Vis-NIR spectroscopy, it is necessary to improve the precision and the robustness of the model for practice.
Prediction of the Amino Acid Composition in Brown Rice Using Different Sample Status by Near-Infrared Reflectance Spectroscopy

Abstract:In this study, 279 samples of brown rice grains and their flour, selected from a larger original population, were scanned by NIRSystem model 5000 mono-chromator in these two kinds of sample status for near-infrared reflectance spectroscopy (NIRS) analysis. Spectral pretreatment method 2,8,8,1 combined with SNV+D scatter correction was found suitable for developing calibration equations for amino acids. Equations for total amino acid content and for all individual amino acids, excluding cystine, methionine and tyrosine, were developed with this spectral pretreatment method. These equations had low SECV (0.010–0.063%) and SEP (0.011–0.066%); with high 1−VR (0.878–0.960), R2 (0.837–0.947) and SD/SEP (2.421–4.333). The results suggest that equations for the thirteen amino acids from the two sample categories can be directly used to estimate the amino acid composition in brown rice. This indicates once more that NIRS is a powerful technology that could be very useful for the determination of amino acid content in breeding programs that involve brown rice as well as for quality control in the food industry.
Qualitative and Quantitative Detection of Minced Pork Quality by Near Infrared Reflectance Spectroscopy

Abstract:The present study is concerning qualitative and quantitative detection of minced pork quality based on FT-near infrared (FT-NIR) spectroscopy and achieving the rapid approach to detecting the minced pork quality. Firstly, FT-NIR spectroscopy combined with partial least squares (PLS) and least squares-support vector machine (LS-SVM) was used for minced pork quality prediction including discrimination of the different muscle type of pig and quantitative detection of the fat, protein and moisture content of pork. The result indicated that 100% recognition ratio for calibration and 96% recognition ratio for validation were achieved by PLSDA for 4 different muscle types of pig. These two methods for chemical composition detection both have good performances in predicting fat and moisture content, the correlation coefficient for calibration and validation was all more than 0.9, but the models for protein content prediction were of less well performances, the correlation coefficients for calibration and validation, RMSEC, RMSEP and RMSECV respectively were 0.722, 0.593, 1.595, 1.550 and 1.888, respectively. The LS-SVM method is more accurate in predicting each quality index than the PLSR method. The result shows that the prediction models for fat and moisture content based on LS-SVM have a better performance with high precision, good stability and adaptability and can be used to predict the fat and moisture content of minced pork rapidly, and provide a fast approach to discrimination of the different muscle type of pig.

Abstract:An electronic nose (e-nose) instrument combined with chemometrics was used to predict the physical–chemical indexes (sensory scores, total volatile basic nitrogen (TVBN) and microbial population) for beef. The e-nose data generated were analyzed by chemometrics methods and pattern recognition. Mahalanobis Distance (MD) analysis, Principle Component Analysis (PCA) and Linear Discriminant Analysis (LDA) conﬁrmed the difference in volatile proﬁles of beef samples of 7 different storage times (ST). The Back Propagation Neural Network (BPNN) and Generalized Regression Neural Network (GRNN) were used to build prediction models for ST, TVBN content, microbial population and sensory scores. The result of GRNN was better than that of BPNN, and the standard error (SE) of GRNN prediction model for ST, TVBN, microbial population, sensory scores were 1.36 days, 4.64×10−2mgg−1, 1.612×106cfug−1 and 1.31 respectively. This research indicates that it is of feasibility to use e-nose to predict multiple freshness indexes for beef.
Non-destructive determination of beef freshness based on colorimetric sensor array and multivariate analysis

Abstract:Rapid and reliable detection of beef freshness is essential for diet safety and resource-saving. In this study, the colorimetric sensor array (CSA) integrated with whale optimization algorithm (WOA) and back-propagation neural network (BPNN) had been innovatively developed for the quantitative determination of beef freshness, regarding the total volatile basic nitrogen (TVB-N) and total viable counts (TVC) contents. Firstly, the CSA comprising twelve color-sensitive dyes was designed to acquire the scent fingerprints (RGB triplets) during beef storage. Secondly, WOA-BPNN was used to optimize the color components combination from the preprocessed CSA to acquire the dominant color components. Finally, the BPNN models were constructed based on the optimized color components, with the BPNN topology of 8-12-1 for TVB-N prediction and 6-6-1 for TVC prediction. The results revealed that the BPNN model combined with optimized color components could be utilized to quantitatively determine beef freshness. The overall results demonstrated that the CSA integrated with appropriate multivariable analysis methods could realize rapid and reliable quantitative determination of beef freshness. Furthermore, the WOA-BPNN could effectively extract the dominant color components, which was beneficial for improving detection accuracy and robustness of the BPNN, as well as time-and cost-saving.

Abstract:Colorimetric sensor array (CSA) and bionic algorithms were integrated to form a facile platform for total volatile basic nitrogen (TVB-N) determination. First, a CSA containing twelve color-sensitive materials was prepared to obtain scent information of beef and generate scent fingerprints for visualization. Second, four bionic optimization algorithms, ant colony optimization (ACO), particle swarm optimization (PSO), simulated annealing (SA), and whale optimization algorithm (WOA), were used to extract the characteristic fingerprint variables from the CSA. Finally, the back-propagation neural network (BPNN) model combined with characteristic color components was constructed to determine the TVB-N during beef storage, with improved precision, robustness, and generalization performance. The results demonstrated that WOA had the best optimization performance, followed by PSO, ACO, and SA. The WOA-BPNN optimized only two materials to detect TVB-N during beef storage. The BPNN constructed by three variables from the two selected materials had the best determination results, with the RMSEC, Rc , RMSEP, Rp , and RPD were 2.502 ± 0.083 mg/100g, 0.966 ± 0.002, 2.903 ± 0.143 mg/100g, 0.952 ± 0.006, and 3.430 ± 0.185, respectively. Therefore, the WOA-BPNN model could realize high-precision quantitative determination of TVB-N during beef storage and save resources for CSA preparation. The combination of CSA and the excellent bionic algorithm is expected to become a facile on-site sensing platform for food freshness monitoring.

Key Variables Screening of Near-Infrared Models for Simultaneous Determination of Quality Parameters in Traditional Chinese Food “Fuzhu”

Abstract:The traditional Chinese food Fuzhu is a dried soy protein-lipid film formed during the heating of soymilk. This study investigates whether a simple and accurate model can nondestructively determine the quality parameters of intact Fuzhu. The diffused reflectance spectra (1000–2499 nm) of intact Fuzhu were collected by a commercial near-infrared (NIR) spectrometer. Among various preprocessing methods, the derivative by wavelet transform method optimally enhanced the characteristic signals of Fuzhu spectra. Uninformative variable elimination based on Monte Carlo (MC-UVE), random frog (RF), and competitive adaptive reweighted sampling (CARS) were proposed to select key variables for partial least squares (PLS) calculation. The strong performance of the developed models is attributed to the high ratios of prediction to deviation values (3.32–3.51 for protein, 3.62–3.89 for lipid, and 4.27–4.55 for moisture). The prediction set was used to assess the performances of the best models of protein (CARS-PLS), lipid (RF-PLS), and moisture (CARS-PLS), which resulted in greater coefficients of determination of 0.958, 0.966, and 0.976, respectively, and lower root mean square errors of prediction of 0.656%, 0.442%, and 0.123%, respectively. Combined with chemometrics methods, the NIR technique is promising for simultaneous testing of quality parameters of intact Fuzhu.

Abstract:The potential of near infrared (NIR) spectroscopy for non-destructive determination of quality parameters including oil and protein contents in shell-intact cottonseed was investigated. Linear partial least squares (PLS) and nonlinear least-squares support vector machine (LS-SVM) methods were used to develop the calibration models to determinate the protein and oil contents. Moreover, as variable selection techniques, the Monte Carlo uninformative variable elimination (MC-UVE) and the successive projections algorithm (SPA) were applied to improve the predictive ability of the model. Finally, the MC-UVE-LS-SVM models show the best prediction performance. The coefficient of determination (R-2), residual predictive deviation (RPD) and root mean squares error of prediction (RMSEP) were 0.959, 4.871 and 0.977 for protein, and 0.950, 4.429 and 0.834 for oil, respectively. The results indicate that NIR technology could be very useful for the rapid quality analysis of shell-intact cottonseed avoiding the need of grinding. Furthermore, the variable selection of MC-UVE can provide more robust and accurate calibration models than SPA. (C) 2012 Elsevier B.V. All rights reserved.

Abstract:Beef is easily spoiled, resulting in foodborne illness and high societal costs. This study proposed a novel olfactory visualization system based on colorimetric sensor array and chemometric methods to detect beef freshness. First, twelve color-sensitive materials were immobilized on a hydrophobic platform to acquire scent information of beef samples according to solvatochromic effects. Second, machine vision algorithms were used to extract the scent fingerprints, and principal component analysis (PCA) was employed to compress the feature dimensions of the fingerprints. Finally, four qualitative models, k-nearest neighbor, extreme learning machine, support vector machine (SVM), and random forest, were constructed to evaluate the beef freshness according to the value of total volatile basic nitrogen (TVB-N) and total viable counts (TVC). Results demonstrated that SVM had a preferable prediction ability, with 95.83% and 95.00% precision in the training and prediction sets, respectively. The results revealed that the simple constructed olfactory visualization sensor system could rapidly, robustly, and accurately assess beef freshness.
Application of Near Infrared Spectroscopy Combined with Particle Swarm Optimization Based Least Square Support Vactor Machine to Rapid Quantitative Analysis of Corni Fructus

Abstract:A novel method was developed for the rapid determination of multi-indicators in corni fructus by means of near infrared (NIR) spectroscopy. Particle swarm optimization (PSO) based least squares support vector machine was investigated to increase the levels of quality control. The calibration models of moisture, extractum, morroniside and loganin were established using the PSO-LS-SVM algorithm. The performance of PSO-LS-SVM models was compared with partial least squares regression (PLSR) and back propagation artificial neural network (BP-ANN). The calibration and validation results of PSO-LS-SVM were superior to both PLS and BP-ANN. For PSO-LS-SVM models, the correlation coefficients (r) of calibrations were all above 0.942. The optimal prediction results were also achieved by PSO-LS-SVM models with the RMSEP (root mean square error of prediction) and RSEP (relative standard errors of prediction) less than 1.176 and 15.5% respectively. The results suggest that PSO-LS-SVM algorithm has a good model performance and high prediction accuracy. NIR has a potential value for rapid determination of multi-indicators in Corni Fructus.
Combination of Spectral and Textural Information of Hyperspectral Imaging for the Prediction of the Moisture Content and Storage Time of Cooked Beef

Abstract:The feasibility of combining spectral and textural information from hyperspectral imaging to predict the moisture content and storage time of cooked beef was explored. A total of 10 optimal wavelengths were selected for the moisture content and storage time by conducting variable combination population analysis (VCPA). Principal component analysis was employed to reduce the number of dimensions of hyperspectral images, while a discrete cosine transform was applied to the first three principal component images to extract 30 textural features. A back-propagation artificial neural network (BP-ANN) model and partial least-squares regression model were developed to predict the moisture content and storage time from spectra, textural data, and their combination. The fused BP-ANN model provided satisfactory results with Rp2 of 0.977, and RMSEP of 0.9151 for the prediction of moisture content; these results were superior to those obtained with spectral or textual information alone. Combined with the storage time, the distribution map of the moisture content of cooked beef was visualized using the best fused BP-ANN model with imaging process method. The results reveal that the combination of spectral and textural information of hyperspectral imaging coupled with the BP-ANN algorithm has strong potential for the prediction and visualization of the moisture content of cooked beef at different storage times.
Application of Electronic Nose and Neural Network in Beef Freshness Detection

Abstract:Fresh beef under 0~12 day cold storage were detected by sensory evaluation, semi-micro determination of nitrogen detection, microbiological testing and electronic nose(e-nose) detection. For the e-nose detection, the 50th s sensor signals were extracted for analysis. Mahalanobis Distance(MD) between fresh and stored samples enlarged with the increase of storage time, and the quality of beef significantly changed after stored for 5 days. Principle component analysis(PCA) and Linear Discriminant Analysis(LDA) results indicated that all the beef samples could be well distinguished except a little overlap between the samples stored for 0~5 days. Stepwise Linear Discriminant Analysis(Step-LDA) was applied to predict the storage time and got an accuracy of 96.19%. Back Propagation Neural Network(BPNN)and Generalized Regression Neural Network(GRNN) were also used to build a correlation model between the storage time and the physicochemical indicators, which showed that GRNN was better than BPNN. The prediction error based on the GRNN model for the storage time, total volatile basic nitrogen, microbial population and sensory scores were 1.36 days, 4.64?10-2 mg/g, 1.61×106 cfu/g and 1.31, respectively.
Rapid Detection of Total Viable Count in Intact Beef Dishes Based on NIR Hyperspectral Hybrid Model

Abstract:The total viable count (TVC) of bacteria is an important index to evaluate the freshness and safety of dishes. To improve the accuracy and robustness of spectroscopic detection of total viable bacteria count in a complex system, a new method based on a near-infrared (NIR) hyperspectral hybrid model and Support Vector Machine (SVM) algorithms was developed to directly determine the total viable count in intact beef dish samples in this study. Diffuse reflectance data of intact and crushed samples were tested by NIR hyperspectral and processed using Multiplicative Scattering Correction (MSC) and Competitive Adaptive Reweighted Sampling (CARS). Kennard-Stone (KS) and Samples Set Partitioning Based on Joint X-Y Distance (SPXY) algorithms were used to select the optimal number of standard samples transferred by the model combined with root mean square error. The crushed samples were transferred into the complete samples prediction model through the Direct Standardization (DS) algorithm. The spectral hybrid model of crushed samples and full samples was established. The results showed that the Determination Coefficient of Calibration (RP2) value of the total samples prediction set increased from 0.5088 to 0.8068, and the value of the Root Mean Square Error of Prediction (RMSEP) decreased from 0.2454 to 0.1691 log10 CFU/g. After establishing the hybrid model, the RMSEP value decreased by 9.23% more than before, and the values of Relative Percent Deviation (RPD) and Reaction Error Relation (RER) increased by 12.12% and 10.09, respectively. The results of this study showed that TVC instewed beef samples can be non-destructively determined based on the DS model transfer method combined with the hybrid model strategy. This study provided a reference for solving the problem of poor accuracy and reliability of prediction models in heterogeneous samples.

Abstract:Rapid non-destructive testing technologies are effectively used to analyze and evaluate the linoleic acid content while processing fresh meat products. In current study, hyperspectral imaging (HSI) technology was combined with deep learning optimization algorithm to model and analyze the linoleic acid content in 252 mixed red meat samples. A comparative study was conducted by experimenting mixed sample data preprocessing methods and feature wavelength extraction methods depending on the distribution of linoleic acid content. Initially, convolutional neural network Bi-directional long short-term memory (CNN-Bi-LSTM) model was constructed to reduce the loss of the fully connected layer extracted feature information and optimize the prediction effect. In addition, the prediction process of overfitting phenomenon in the CNN-Bi-LSTM model was also targeted. The Bayesian-CNN-Bi-LSTM (Bayes-CNN-Bi-LSTM) model was proposed to improve the linoleic acid prediction in red meat through iterative optimization of Gaussian process acceleration function. Results showed that best preprocessing effect was achieved by using the detrending algorithm, while 11 feature wavelengths extracted by variable combination population analysis (VCPA) method effectively contained characteristic group information of linoleic acid. The Bi-directional LSTM (Bi-LSTM) model combined with the feature extraction data set of VCPA method predicted 0.860 Rp2 value of linoleic acid content in red meat. The CNN-Bi-LSTM model achieved an Rp2 of 0.889, and the optimized Bayes-CNN-Bi-LSTM model was constructed to achieve the best prediction with an Rp2 of 0.909. This study provided a reference for the rapid synchronous detection of mixed sample indicators, and a theoretical basis for the development of hyperspectral on-line detection equipment.
Combining Vis-NIR and NIR hyperspectral imaging techniques with a data fusion strategy for the rapid qualitative evaluation of multiple qualities in chicken

Abstract:Total volatile basic nitrogen (TVB-N) and total viable count (TVC) are two important indicators for evaluating and controlling the quality and safety of chicken fillets. The aim of this study is to evaluate two hyperspectral imaging techniques (visible near-infrared (Vis-NIR) and NIR) in combination with low-level and intermediate-level fusion strategies (LLF and ILF) for the prediction of multiple quality indicators of chicken fillets stored at 4 °C. Quantitative predictions using partial least squares regression (PLSR) were established after preprocessing and feature wavelength selection. The results showed that the data fusion strategy exhibited better performance in both indicators compared to individual data. The LLF strategy showed optimal performance in predicting the TVC content with an RP2 of 0.9275 and an RMSEP of 0.1889, while the ILF strategy was best in predicting the TVB-N content with an RP2 of 0.8652 and an RMSEP of 2.6094. Moreover, the optimal models based on selected bands were used to achieve visual maps of the TVB-N and TVC contents. Although validation with an independent batch of samples was not used, it was a feasibility and valuable study. The experiment results demonstrated that the fusion of two types of hyperspectral data can be successfully used to evaluation of chicken multiple qualities, and provided a potential method for monitoring and detection of meat qualities.

A pH-Responsive colourimetric sensor array based on machine learning for real-time monitoring of beef freshness

Abstract:A novel strategy based on a pH-responded colourimetric sensor array (CSA) was developed by combining it with machine learning models to effectively monitor the freshness of beef in real time through the detection of total volatile basic nitrogen (TVB-N) contents. A total of 168 colour features were calculated and effective colour features sensitive to the changes in TVB-N contents were extracted by sequential forward selection (SFS), random forest (RF), and principal component analysis (PCA). Besides, the linear regression model of partial least squares regression (PLSR) as well as nonlinear regression models of random forest regression (RFR) and support vector machine regression (SVR) were established to predict TVB-N values of beef at 28 °C based on full and effective colour features. The RF-SVR model had the best performance with a corresponding determination coefficient of prediction (R p 2 ) of 0.9596, a root-mean-square error of prediction (RMSEP) of 1.89 mg/100 g, and a relative prediction deviation (RPD) of 4.98. Moreover, the CSA based on the RF-SVR model was applied to the quantitative analysis of beef freshness at 4 °C storage, validated by using a standard method for the detection of TVB-N contents in beef samples. The results illustrated that the CSA as an objective and nondestructive tool can monitor TVB-N contents for the evaluation of beef freshness with the help of machine learning.

Abstract:Electrical impedance spectroscopy (EIS) combined with machine learning is a popular method for meat quality inspection. However, EIS data is sensitive to temperature fluctuations, necessitating a waiting period under stable temperature conditions for data stabilisation. To address this, standardisation, normalisation, and smoothing techniques were introduced to EIS data. This study shows that consistent temperature conditions are not necessary when proper spectra pre‐processing methods are applied. Summary The fraudulent practice of beef adulteration is a growing concern, as it violates consumer rights. Electrical impedance spectroscopy (EIS) combined with machine learning has emerged as a widely used approach to identify low‐quality meat. Unlike traditional biochemical methods that require expensive instruments, complex sample preparation, and chemical reagents, EIS is a cost‐effective alternative. However, EIS data are susceptible to temperature fluctuations, requiring a waiting period under consistent temperature conditions for data stabilisation before measurements. This process becomes impractical when dealing with a large number of samples. To overcome this limitation, standardisation, normalisation, and smoothing methods were introduced in the meat quality detection based on EIS data. A recognition model for detecting carrageenan adulteration in beef was established. Under an inconsistent temperature condition, by applying the spectra pre‐processing methods to the prediction dataset, the model accuracy reached 84%, whereas the accuracy of the unprocessed prediction dataset dropped to 54%. This study demonstrates that acquiring EIS data under consistent temperature conditions is unnecessary if proper spectra pre‐processing methods are applied. By eliminating the waiting time for data stabilisation, this practical approach enhances the efficiency and accuracy of meat quality detection.
