Abstract:Robot calibration is used to improve the accuracy of the kinematic model to achieve the higher positioning accuracy within the workspace. Due to some nongeometrical reasons such as joint and link flexibility, the errors are unevenly distributed in the workspace. In this case, it is difficult for the existing methods used to improve the absolute positioning accuracy to achieve good results in each region, especially for robots with large self-weights. In this paper, a novel calibration method is proposed, which deals with joint deflection dependent errors to enhance the robot positioning accuracy in the whole workspace. Firstly, the joint angle workspace is divided into several local regions according to the mass distribution of the robot. Then, its geometric parameters are modeled and identified using the Denavit–Hartenberg (DH) model in each region and in the whole workspace separately. Since the nongeometric error sources are difficult to model correctly, an artificial neural network (ANN) is applied to compensate for the nongeometric errors. Finally, the experiments using an 8 degree-of-freedom (DOF) engineering robot are conducted to demonstrate the validity of the proposed method. The combination of the joint angle division and ANN could be an effective solution for the robot calibration, especially for one with a large self-weight.
An Efficient Temperature Calibration Method Based on the Improved Infrared Forward Model and Bayesian Inference

Abstract:Infrared thermography is widely used to detect abnormal body temperature because of its noncontact and large scale. Attenuation during infrared propagation causes the measured temperature to always be less than the actual value. This article proposes a novel method of temperature calibration based on Bayesian inference. In the first step, we propose an improved infrared radiation model (IIRM), which accounts for emissivity and measures the distance between the radiation source and the infrared imager. This study leverages naive Bayesian inference (NBI) to derive surface emissivity. Then, using the improved model, the parameters of the model and the temperature distribution are reconstructed by joint maximum a posterior (JMAP). The IIRM and JMAP method (IIRM-JMAP) improved the accuracy of temperature measurement. The improved infrared thermal radiation model is suitable for measuring scenarios with different measuring distances, different humidity factors, and different emissivities. The proposed method has been validated to have small errors through various experiments on a blackbody and high-speed direct-drive blower.

Abstract:Background: A thermistor is a nonlinear sensor requiring a precise calibration technique to achieve accurate temperature measurements. This paper attempts to design a calibration technique employing artificial neural network (ANN) algorithms. The present work fulfills the following objectives: (i) to cover 100% input range in the linearity range measurement; (ii) to make the measurement technique adaptive to variations in reference resistance and thermistor temperature coefficient using a calibration technique. Methods: An ANN-based calibration circuit is cascaded to the data conversion circuit. Optimized ANN is trained with linear data independent of reference resistance and temperature coefficient effects on thermistor output. ANN optimization is performed by comparing various schemes, algorithms, and numbers of hidden layers to achieve a minimum mean square error and a regression close to 1. Results: The proposed technique provides a linear relationship for the system over the entire input range and avoids the requirement of repeated calibrations each time the thermistor is replaced. Practical data are used to validate the proposed measurement technique. Conclusions: The objectives and proposed technique have been demonstrated by results with a root mean square percentage error of 1.8%.

Development of an Automatic Calibration Device for High-Accuracy Low Temperature Thermometers

Abstract:Based on the analysis and investigation of calibration systems for high-accuracy low temperature thermometers, a new facility for automatic calibration of high-accuracy low temperature thermometers was developed. Continuous calibration for multiple points can be made automatically with this device. According to the thermophysical characteristics of the constant-temperature block in this device, segmented Fuzzy-PID (proportional-integral-differential) algorithm was applied. The experimental results showed that the temperature fluctuation was smaller than ±0.005 K in 30 min. Therefore, this new device can fully meet the calibration requirement of high-precision low temperature thermometers.

Abstract:Urban air quality information, e.g., PM2.5 concentration, is of great importance to both the government and society. Recently, there is a growing interest in developing low-cost sensors, installed on moving vehicles, for fine-grained air quality measurement. However, low-cost mobile sensors typically suffer from low accuracy and thus need careful calibration to preserve a high measurement quality. In this paper, we propose a two-phase data calibration method consisting of a linear part and a nonlinear part. We use MLS (multiple least square) to train the linear part, and use RF (random forest) to train the nonlinear part. We propose an automatic feature selection algorithm based on AIC (Akaike information criterion) for the linear model, which helps avoid overfitting due to the inclusion of inappropriate features. We evaluate our method extensively. Results show that our method outperforms existing approaches, achieving an overall accuracy improvement of 16.4% in terms of PM2.5 levels compared with state-of-the-art approach.

Abstract:A novel method based on Least Square Support Vector Machine(LS-SVM) and genetic algorithm to select the temperature sensors of a Numerical Control(NC) machine tool was presented.The measurement points in a CNC lathe were grouped based on the thermal mode theory,Then,the genetic algorithm was used to determine the positions of optimum sensors.Finally,a thermal error regression model was established by the LS-SVM and a compensation model for the machine tool was given also.The results show that the novel method combined genetic algorithms and LS-SVM well avoids the correlation of the temperature sensors and ensures the accuracy of the model.In the experiments of the CNC lathe,the mean Absolute percentage error of the LS-SVM model is 1.89% in axial direction and 2.04% in radial direction,it also can reduce costs and shorten modeling time for less temperature sensors.
A Soft Calibration Technique for Infrared Imaging Based on Physical Model of Thermal Radiation and Variational Bayesian Inference from Small Dataset

Abstract:Nowadays, infrared thermal imaging has been widely used as a non-contact, long-distance, and large-scale temperature measurement method. Nonetheless, the temperature measurement process of the infrared sensor is affected by several factors, such as the measurement distance, the emissivity of the object’s surface, the ambient temperature, and so on. Therefore, there is still considerable error between the measured temperature and the ground-truth one. Two significant factors severely limit the temperature calibration: the complex factors mentioned above and the lack of big data for learning nonlinear-mapping. This paper proposes a soft-calibration approach of infrared imaging temperature based upon the combination of the physical model of thermal radiation (PMTR) and variational Bayesian inference (VBI). Rather than big-data mining, the proposed method can combine PMTR and the sparsity-enforcing prior of the infrared image, therefore using the VBI algorithm to learn the nonlinear mapping relationships from a limited dataset. Moreover, the exponential potential prior is properly assigned to the Bayesian inference process and the Kullback-Leibler (KL) divergence criterion is adopted for the optimization process. The soft calibration of a cost-effective of infrared sensor has been carried out through the experiment. The result shows that the temperature calibration errors of our method are within $1.0 ^{\circ}\mathrm{C}$, which is better than the Maximum A Posterior (MAP) method, the artificial neural network (ANN) method, and so on.

Abstract:Nonlinear error compensation is a significant factor that affects the measurement accuracy of temperature sensors. Cryogenic temperature sensors require a precise calibration technique to achieve accurate temperature measurements. BP (Back Propagation) neural networks are not suitable for sensor temperature prediction due to slow convergence and poor learning ability. In this study, a Chebyshev polynomial-based BiLSTM (Bi-directional Long Short-Term Memory) algorithm (C-BiLSTM) is proposed to improve the accuracy of measurement. Firstly, we demonstrate vacuum packaged temperature sensors based on zirconium oxynitride (ZrO x N y ) thin films with ultra-high sensitivity at cryogenic temperatures. Secondly, a dataset consisting of sensor resistance and temperature values was obtained from five above-mentioned sensors, which contains 29 calibration points in the temperature range of 16 K-300 K measured by the Calibration System. Then, the dataset was divided into two temperature ranges (16 K-54.358 K and 40 K-300 K). In the range 16–54.358 K, 14 set-points are selected as training set and 3 set-points as testing set. In the range 40–300 K, 12 set-points are selected as training set and 2 set-points as testing set. Thirdly, a neural network model was built and trained using the TensorFlow framework. By comparing C-BiLSTM we proposed with the BP neural network and BiLSTM, the results show that the C-BiLSTM model converges faster and greatly improves the prediction accuracy after adding Chebyshev polynomial features. The fitting error and prediction error are less than 1 mK in the temperature range of 16 K-40 K. They can also keep less than 10 mK even at the wide temperature range of 40 K-300 K, which is a significant improvement respect to improving the accuracy of temperature measurement.

Abstract:This paper introduces a novel sensor calibration scheme, the Hybrid Analytical and Network (HAN) model, which is especially suitable for regression based on neural networks with small training datasets. Through the HAN model, qualitative physical knowledge can be used to facilitate network training so that the demand on training data can be significantly reduced. Furthermore, training results can be transferred to the calibration of other types of sensors. The HAN model has been used to calibrate two haptic sensors, namely, the balance sensor and the skin sensor, which both operate on the principle of Frustrated Total Internal Reflection (FTIR), but for two different applications. The balance sensor is designed for human balance ability assessment, while the skin sensor is designed for evaluation of human skin properties. The calibration results using the HAN model are far more accurate and faster than other neural network training methods, especially for a small experiment dataset. The strong transfer ability of the HAN model is also demonstrated by the transfer attempt from balance sensor calibration to that of the skin sensor. The HAN model provides a new method to integrate model-based and data-driven sensor calibration methods, and shows greater efficacy. Its application is not restricted to sensor calibration but has broader potential value in all neural network regression tasks.

Abstract:Thermal errors account for a significant part of the dimensional errors of components produced by precision machine tools. These errors are commonly compensated using predictions from temperature-based empirical models. The accuracy and robustness of these predictions are affected by the locations of temperature sensors used to obtain the model's input data. Methods for sensor selection found in literature are often difficult to replicate and automate because they require tuning of several hyperparameters. This work presents a sensor and model selection approach that uses proper orthogonal decomposition (POD) and QR pivoting to select a subset of sensors that have been preinstalled in the machine tool as possible model inputs. These sensors are then sorted according to their correlation with the thermal error being modelled. The final set of inputs and thermal error model structure is chosen using Bayesian Information Criterion (BIC) to limit model overfitting. The approach was tested by modelling the Y -axis thermal error measured from air-cutting experiments performed under different spindle speeds and feed rates. This enabled determination of the structure and the choice inputs for Adaptive Neuro Fuzzy Inference System (ANFIS) and Artificial Neural Network (ANN) thermal error models. The accuracy of these models was compared to that of models trained using inputs selected by conventional approaches: the least absolute shrinkage and selection operator (LASSO), fuzzy c-means clustering (FCM), and principal component regression (PCR). The presented approach had better or comparable results to the conventional approaches while using fewer inputs. The presented approach is also well suited for automation compared to conventional approaches that require expert input.

Abstract:Continuous body temperature measurement (CBTM) is of great significance for human health state monitoring. To avoid interfering with users daily activities, CBTM is usually achieved using wearable noninvasive thermometers. Current wearable noninvasive thermometers employ steady-state models used in nonwearable thermometers; as a result, the reaction time is long and the measurement can be disturbed by users activities. However, there is no work to solve these issues. In this paper, first, differences between wearable and nonwearable temperature measurement are analyzed. Second, the relationship among the human body temperature, the skin temperature, and the device temperature is modeled based on artificial neural networks (ANNs). Third, this paper proposes a novel multiple ANNs-based wearable CBTM method. Experiments show that the reaction time of the proposed method is about one-tenth of that of other popular wearable noninvasive CBTM methods, while the accuracy and the robustness are improved.

Assessment and Calibration on Low-cost PM2.5 Sensor using Machin Learning (Hybrid-LSTM Neural Network): Feasibility Study to Build Air Quality Monitoring System

Abstract:Although commercially-available low-cost air quality sensors have low accuracy, the sensor system are being used to collect the data for the regulation of PM2.5 emission caused by industrial activities or to estimate the personal exposure for PM2.5. In this work, to solve the accuracy problem of low-cost PM sensor, we developed a new PM2.5 calibration model by combining the deep neural network (DNN) optimized in calibration problem and a LSTM optimized in time-dependent characteristics. First, two datasets were generated to test the accuracy performance and generalization performance of the PM2.5 calibration machine learning (ML) model. The PM2.5 concentrations, temperature and humidity by low-cost sensor and gravimetric-based PM2.5 measuring instrument were sampled for a sufficiently long time. The proposed model was compared with benchmark (multiple linear regression model) and low-cost sensor results. For root mean square error (RMSE) for PM2.5 concentrations, the proposed model reduced 41-60% of error compared to the raw data of low-cost sensor, and reduced 30-51% of error compared to the benchmark model. R2 of ML model, MLR and raw data were 93, 80 and 59 %. Also, the developed model still showed consistent calibration performance when calibrated with new sensors in different locations. Low-cost sensors combined with ML model not only can improve the calibration performance of benchmark, but also can be applied to the sensor monitoring systems for various epidemiologic investigations and regulatory decisions.
Machine learning-based predictive model for temperature and comfort parameters in indoor enviroment using experimantal data

Abstract:The research introduces an artificial neural network model that predicts temperature and assesses thermal comfort metrics for a cooling room, demonstrating how machine learning advancements can enhance thermal efficiency and cost-effectiveness in building design. The study utilized the Levenberg-Marquardt (LM) artificial neural network (ANN) approach to derive the average temperature and thermal comfort metrics collected under actual operating settings. The Predicted Mean Vote (PMV) and Predicted Percentage Dissatisfied (PPD)values were measured at three distinct sites and then compared to the trial findings. The model uses a dataset of 205 observations, with 143 cases used for training and 31 examples for testing and validation. The ANN model demonstrated effective training, with negligible errors in estimated error values. The mean squared error values for average temperature and thermal comfort parameters were 0.0342, 0.0376, 0.0571, 0.0029, and 0.2296. The R values for temperature measurements are 0.9947 and 0.9923, 0.9847 and 0.9437, and 0.9737, demonstrating a highly effective engineering method. The ANN model provided precise predictions for temperature and thermal comfort metrics, such as PMV and PPD in a cooling chamber, with a tolerance of ± 15 %. The LM approach, a machine learning methodology, produced excellent outcomes, particularly at lower temperatures, with 15 % of the data exceeding this range.

Research of neural network-based model for nonlinear temperature drift compensation of MEMS accelerometers

Abstract:Downhole instrumentation requires more and more accuracy of MEMS inertial sensors. However, in measurement while drilling, temperature drift phenomenon of the sensor will have a cumulative impact on the drill pipe attitude solution. After experimental testing, the output response of the accelerometer had strong local linear and global nonlinear characteristics. In this paper, we proposed a temperature compensation model based on tent chaotic mapping and sparrow search algorithm optimized back propagation (BP) neural network (Tent-SSA-BPNN). Sparrow search algorithm (SSA) was optimized by tent chaotic mapping, which was utilized to improve the uniformity and search ability of SSA populations. Then, the improved SSA was used to optimize the weight and bias parameters of the BP neural network for constructing the temperature compensation model. Finally, the trained compensation model is integrated into the microprogram control unit for real-time compensation testing. The experimental results show that after sacrificing a small amount of sampling frequency, the compensation model proposed in this article has good global compensation performance, and the mean absolute percentage error is reduced from 2% to 0.2% compared to the original output. The mean absolute error and root mean square error of the improved compensation model are all reduced compared to the pre-improved BP compensation model. This temperature-compensated modeling method has a reference value for low-cost and high-precision modeling in high temperature environments, while greatly saving time cost and measurement costs.

Abstract:In this article, we present the statistical analysis of data from inexpensive sensors. We also present the performance of machine learning algorithms when used for automatic calibration of such sensors. In this, we have used low-cost nondispersive infrared CO2 sensor placed at a co-located site at Cape Point, South Africa (maintained by Weather South Africa). The collected low-cost sensor data and site truth data are investigated and compared. We compare and investigate the performance of random forest regression, support vector regression, 1-D convolutional neural network (CNN), and 1D-CNN long short-term memory network models as a method for automatic calibration and the statistical properties of these model predictions. In addition, we also investigate the drift in performance of these algorithms with time.

Field-aware Calibration: A Simple and Empirically Strong Method for Reliable Probabilistic Predictions

Abstract:It is often observed that the probabilistic predictions given by a machine learning model can disagree with averaged actual outcomes on specific subsets of data, which is also known as the issue of miscalibration. It is responsible for the unreliability of practical machine learning systems. For example, in online advertising, an ad can receive a click-through rate prediction of 0.1 over some population of users where its actual click rate is 0.15. In such cases, the probabilistic predictions have to be fixed before the system can be deployed. In this paper, we first introduce a new evaluation metric named field-level calibration error that measures the bias in predictions over the sensitive input field that the decision-maker concerns. We show that existing post-hoc calibration methods have limited improvements in the new field-level metric and other non-calibration metrics such as the AUC score. To this end, we propose Neural Calibration, a simple yet powerful post-hoc calibration method that learns to calibrate by making full use of the field-aware information over the validation set. We present extensive experiments on five large-scale datasets. The results showed that Neural Calibration significantly improves against uncalibrated predictions in common metrics such as the negative log-likelihood, Brier score and AUC, as well as the proposed field-level calibration error.
Calibration Furnace Temperature Control System Based on RBF Neural Network

Abstract:In order to improve the control property of the calibration furnace(for thermocouple verification) temperature,studies on method of model on-line identification of calibration furnace based on RBF neural network and self-tuning parameters of the PID controller,designs an intelligent control system about calibration furnace temperature. Since the calibration furnace is a nonlinear and non-stationary complex object. Firstly,using RBF neural network to identify the relationship between the calibration furnace input and output,then,based on the minimum standard deviation,regulates the PID parameters by the method of gradient descent, finally,realize intelligent control of the calibration furnace temperature. The test results show that the controller that based on RBF neural network has better performance in regulating the calibration furnace temperature in the 200 ~ 1 200 ℃ interval than the traditional PID controller,and up to the requirements that about temperature error and temperature fluctuation degree which described in the national standard.

Abstract:Sensor networks are playing an increasingly important role in modern buildings. With the growing size of building sensor networks and the increasing use of low-cost sensors, the accuracy and reliability of these sensor networks face challenges. Therefore, in-situ calibration of sensor networks is crucial to maintain data quality. Various state-of-the-art methods typically require meeting stringent conditions, such as reference sensors or co-located sensors, accurate physical models, and a large amount of operational data, limiting their applicability in some scenarios. This paper addresses a common issue in sensor calibration: the non-differential calibration issue in uncontrolled environments. We propose an in-situ calibration method based on virtual samples and Autoencoder. Virtual samples are generated through Monte Carlo sampling to ensure the completeness of sample information. Autoencoder autonomously establishes relationships within the sensor network, integrating sensor fault detection and calibration into one step. Offline experiments optimize methods, and online experiments are utilized for verification and analysis. The online experiments demonstrated that the proposed method achieved a calibration accuracy above 98.9 % for single and multiple sensor faults, with a calibration error below 3 %. Compared to the SoT methods, our approach consistently delivered superior performance, confirming its outstanding efficacy.

Abstract:Abstract In this paper, we study the post-hoc calibration of modern neural networks, a problem that has drawn a lot of attention in recent years. Despite the plethora of calibration methods proposed, there is no consensus yet on the inherent complexity of the task and, while some authors claim that simple functions solve the problem, others suggest that more expressive models are needed to capture misscalibration. As a first approach, we focus on the task of confidence scaling, specifically on post-hoc methods that generalize Temperature Scaling, which we refer to as the Adaptive Temperature Scaling family. We begin by demonstrating that while complex models like neural networks provide an advantage when there is ample data, they fail in scenarios where it is limited, notably common in fields like medical diagnosis. We then show how under this ideal data conditions the more expressive methods learn a relationship between the entropy of a prediction and its level of overconfidence, and based on this observation, we propose Entropy-based Temperature Scaling, a simple method that scales the confidence of a prediction according to this relationship. Results show that our method obtains state-of-the-art performance and is robust against data scarcity. Moreover, our proposed model enables a deeper understanding of the calibration process by the interpretation of the entropy as a measure of uncertainty in the network outputs.

Abstract:Effective and accurate measurement of cutting temperature of the tool tip is of great significance in the machining fields. However, the current measuring methods, including the embedded thermocouple and thermography, have some inevitable shortages. For example, the hole for displacing the embedded thermocouple damages the cutting edge strength, and the chip blocks the view contact between the tool tip and the thermal imager. This paper proposes two feed-forward multi-layered perceptron artificial neural network (ANN) models with Levenberg-Marquardt backpropagation training algorithms to determine the tool steady-state tip temperature for the dry turning process. The first model (called TC_ANN) calculates the steady-state tip temperature based on the temperatures of four specific points on the rake face. The second model (called TP_ANN) predicts the steady-state tip temperature via the cutting parameters. First, a fully thermo-mechanical finite element simulation model of the dry turning process is established. Next, the simulation model is repeated with different combinations of cutting parameters for sufficient times. Then, collection of the steady-state temperatures of the tool tip and these four specific points, and corresponding cutting parameters for each simulation model is conducted as the dataset to train these two ANN models. Based on the evaluation results with experimental data, the simulation model is validated to be reliable, and the mean relative errors of the tip temperature calculation for the actual turning process via TC_ANN and TP_ANN are 3.25% and 4.03%, respectively. Finally, the influences of cutting parameters on the tool tip temperature are investigated based on TP_ANN. It is found that the cutting speed and depth of cut have the most and least significant effects on the tip temperature, respectively, and the feed rate has almost the same influence as the depth of cut.
