Abstract:Soil is considered the fundamental factor involved in the survival and development of human beings. The risk of heavy metal pollution in soil has been also increasing yearly along with the continuous advancement of industrialization and urbanization in China. In order to study the scientific perspective of heavy metal pollution prediction of site soil based on non-sampling multi-source heterogeneous data as well as exploring the importance and influence rules of different variables in different heavy metal pollution, 104 typical polluted sites in Zhejiang Province have been selected as the research objects. The site soil heavy metal pollution risk identification index system has been constructed based on the principle of mass balance, including four major variables of enterprise production, atmospheric deposition, plant enrichment, and soil leaching along with twenty Secondary variables. Random Forest and Feature Importance analyzing methods have been used to establish prediction models and explore the importance of variables using detailed site soil pollution survey results. The results have shown that:（1） The mean value of the determination coefficient(R mean ~2=0.75) of the prediction model based on the site mean value of Random Forest has been found higher than that of the models based on the site maximum value(R mean ~2=0.62). The predicting ability of the model method towards the mean values of heavy metal pollution in sites has been found better than that of the maximum values in sites. The preciseness of the prediction models based on the mean values has been ranked as nickel, mercury, cadmium, lead, copper and arsenic from high to low, while the rank based on the maximum values is cadmium, nickel, arsenic, lead, copper and mercury from high to low. The determination coefficient of the prediction model based on the Nemerow comprehensive pollution index（R~2=0.84） has been found higher than the average level of the single heavy metal prediction models and lower than the mean-based prediction models of nickel（R~2=0.92） and mercury（R~2=0.91）；（2） The model has shown poor predicting ability for extremely high values, and the multi-source heterogeneous database has shown weak representing ability for such samples, which could be the main reason why the overall accuracy of the model based on the maximum value has been found lower than that of the model based on the mean value；（3）Based on the average importance of the characteristics, the industrial-environmental impact grade（15.57%）, the proportion of soil clay particles（9.55%）, the highway density（8.44%）, the enterprise operation time（7.31%）, the solar radiation intensity（7.06%）, and the enterprise establishment time（6.56%） have been addressed as the variable indicators closely related to soil heavy metal pollution. The purpose of this study has been set to provide a new approach to the analysis of heavy metal pollution in soil, which includes using multi-source heterogeneous data to identify potential areas where heavy metal pollution risks may exist, analyzing the important relationship between different heavy metal elements and feature variables, and providing more accurate information for the investigation of heavy metal pollution in soil and environmental protection.

A Methodological Framework for Identifying Potential Sources of Soil Heavy Metal Pollution Based on Machine Learning: A Case Study in the Yangtze Delta, China

Abstract:It is a great challenge to identify the many and varied sources of soil heavy metal pollution. Often little information is available regarding the anthropogenic factors and enterprises that could potentially pollute soils. In this study we use freely available geographical data from a search engine in conjunction with machine learning methodologies to identify and classify potentially polluting enterprises in the Yangtze Delta, China. The data were classified into 31 separate and four integrated industry types by five different machine learning approaches. Multinomial naive Bayesian (NB) methods achieved an accuracy of 87% and Kappa coefficient of 0.82 and were used to classify the geographic data from more than 260,000 enterprises. The relationship between the different industry classes and measurements of soil cadmium (Cd) and mercury (Hg) concentrations was explored using bivariate local Moran's I analysis. The analysis revealed areas where different industry classes had led to soil pollution. In the case of Cd, elevated concentrations also occurred in some areas because of excessive fertilization and coal mining. This study provides a new approach to investigate the interaction between anthropogenic pollution and natural sources of soil heavy metals to inform pollution control and planning decisions regarding the location of industrial sites.

Abstract:Often available for use, previously developed land, which includes residential and commercial/industrial areas, presents a significant challenge due to the risk to human health. China's 2018 release of health risk assessment standards for land reuse aimed to bridge this gap in soil quality standards. Despite this, the absence of representative indicators strains risk managers economically and operationally. We improved China's land redevelopment approach by leveraging a dataset of 297,275 soil samples from 352 contaminated sites, employing machine learning. Our method incorporating soil quality standards from seven countries to discern patterns for establishing a cost-effective evaluative framework. Our research findings demonstrated that detection costs could be curtailed by 60% while maintaining consistency with international soil standards (prediction accuracy = 90-98%). Our findings deepen insights into soil pollution, proposing a more efficient risk assessment system for land redevelopment, addressing the current dearth of expertise in evaluating land development in China.

Abstract:In real-world scenarios involving groundwater contamination, the environmental complexity substantially complicates the tasks of tracing pollution sources and characterizing the features of affected sites. To address these challenges, this study presents an integrated framework that combines deep learning (AR-Net-DA) with data assimilation (ES-MDA). This approach effectively traces pollution sources and characterizes site features using sparse data from complex contamination scenarios. The paper introduces a case study involving multisource heavy metal (manganese) pollution in the Hun River basin, Liaoning Province, China. A high-fidelity model for groundwater flow and solute transport was developed. Subsequently, the innovative convolutional neural network model, AR-Net-DA, was employed to replace traditional process-based groundwater models by dynamically optimizing weights in proximity to various pollution sources. This model was then integrated into the ES-MDA inversion framework to concurrently determine pollution source parameters and the spatial distribution of aquifer permeability fields. The results demonstrate that this coupled inversion framework can accurately pinpoint pollution source locations and their release histories using limited observational data, while also mapping the spatial distribution of hydraulic conductivity fields with enhanced computational efficiency. These findings have significant implications for groundwater resource management, pollution risk control, and the remediation of contaminated sites.

Abstract:The accurate identification of pollution sources is important for controlling soil pollution. However, the widely used Positive matrix factorization (PMF) model generally relies on knowledge and experience to accurately identify pollution sources; thus, this method faces significant challenges in objectively identifying soil pollution sources. Herein, we established a comprehensive source analysis framework using factor identification and geospatial analysis, and revealed the factors contributing to trace metal(loid) (TM) pollution in soil in the Pearl River Delta (PRD), China. Using the PMF model, we initially considered that the PRD may be affected by natural, atmospheric, traffic and industrial, and agricultural sources. Moreover, Geodetector model detected the relationship between TMs and 12 environmental variables based on the strong spatial “source–sink” relationship of pollutants. The parent material and digital elevation model were the key factors predicting the accumulation of Cr, Ni, and Cu. Industries and roads were the most important determinants of Pb, Zn, and Cd, whereas atmospheric deposition was more important for Hg accumulation. The accumulation of As was found to be closely related to agricultural activities such as the application of chemical fertilizers and pesticides. The spatial autocorrelation between soil TM pollution and environmental variables further supports this hypothesis. Overall, the obtained results showed that proposed approach improved the accuracy of source apportionment and provided a basis for soil pollution control.

Abstract:Conventional methods for identifying soil heavy metal (HM) pollution sources are limited to area scale, failing to accurately pinpoint sources at specific sites due to the spatial heterogeneity of HMs in mining areas. Furthermore, these methods primarily focus on existing solid waste polluted dumps, defined as "direct pollution sources", while neglecting existing HM pollution hotspots generated by historical anthropogenic activities (e.g., mineral development, industrial discharges), defined as "potential pollution sources". Addressing this gap, a novel remote sensing analysis method is proposed to identify both direct and potential pollution sources at site scale, considering source-sink relationships. Direct pollution sources are extracted using a supervised classification algorithm on high-resolution multispectral imagery. Potential pollution sources depend on the spatial distribution of HM pollution, mapped using a machine learning model with hyperspectral imagery. Additionally, a source identification algorithm is developed for gridded pollution source analysis. Validated through a case study in a cadmium (Cd)-polluted mine area, the proposed method successfully extracted 21 solid waste polluted dumps with an overall accuracy approaching 90 % and a Kappa coefficient of 0.80. Simultaneously, 4167 HM pollution hotspots were identified, achieving optimal inversion accuracy for Cd (Rv2 = 0.91, RMSEv = 4.27, and RPDv = 3.02). Notably, the spatial distribution patterns of these identified sources exhibited a high degree of similarity. Further analysis employing the identification algorithm indicated that 3 polluted dumps and 258 pollution hotspots were pollution sources for a selected high-value point of Cd content. This innovative method provides a valuable methodological reference for precise prevention and control of soil HM pollution.

Abstract:The efficacy of source apportionment is often limited by a lack of information on natural and anthropogenic contributing factors influencing soil heavy metal (HM) contaminations. To overcome this limitation and develop the data mining methods, a novel hybrid data-driven framework was proposed to diagnose the contributing factors in an industrialized region in Guangdong Province, China, mainly using a combination of naive Bayes (NB), random forest (RF), and bivariate local Moran’s I (BLMI) on the basis of the multi-source big data. The medium industry types of enterprises from the freely available Baidu point of interest data were successfully classified, and then the 250 contaminating enterprises as a contributing factor were identified by the optimized NB classifier. The quantitative contributions of the nine contributing factors for the As, Cd, and Hg concentrations were determined by the optimized RF. The twelve spatial clustering maps between the three HM concentrations and the four key contributing factors were generated by BLMI, explicitly revealing their mutual interactions and internal effects and also intuitively showing the “high-high” areas and their distributions. This framework can obtain rich information on contributing factors such as medium industry types, contribution rates, spatial clusters, and spatial distributions.

Abstract:Identifying the current pollution status, future trends, and driving factors is a crucial prerequisite for protecting and managing soil environmental quality in light of the challenging soil heavy metal pollution situation. In this study, a typical industrial city in southeast China was selected as the study area. The environmental capacity of 12 heavy metals was first measured for the evaluation of soil heavy metal pollution, and then spatiotemporal change was simulated using indicator Kriging to warn the pollution risk. Finally, the driving factors of heavy metal pollution were analyzed using random forest and geographical detectors. The results revealed that the average environmental capacity index was 0.768, at a medium capacity level. The environmental capacity of each heavy metal showed a decreasing trend from 2016 to 2035. In 2035, the dynamic environmental capacity of each heavy metal element will have decreased by more than 75% if no preventative and remedial measures are taken. The distance from rivers, fine particulate matter, organic matter content, population density, and distance from industrial enterprises were the main factors contributing to heavy metal pollution in soil. The interaction effect of two environmental factors will mostly lead to the intensification of pollution. Based on the results, this study discussed strategies for controlling and remediating the polluted land. These findings could support the source investigation and early warning of soil heavy metal pollution, which are crucial to manag soil pollution and alleviating environmental quality issues.

Abstract:The intricate and multifaceted nature of soil system profoundly influences the highly complex and often nonlinear changes that soil heavy metals (HM) undergo. Spatial heterogeneity, location and scale variability, and the interaction and superposition among environmental drivers challenged researchers to determine the sophisticated nature of soil HMs changes at the regional scale. This study aims to develop a new method framework and selects Ningbo as the case study to apportion the environmental factors responsible for soil HMs pollution that include Cd, Cr, Pb, Hg, As, Cu, Zn and Ni, focusing on nonlinearity and interaction. We harnessed the Random Forest model to apportion the environmental drivers of soil HM change. The directionality and shape of the nonlinear relationship between HMs and their individual contributors were derived by Partial Dependence Plots. The interactions of multiple drivers were quantitatively assessed by the Conditional Inference Tree. Our results demonstrated that soil HMs in the study area varied spatially. Soil HMs pollution was mitigated by natural factors and anthropogenic factors. The main influencing factors were pH, soil parent material type, enterprise activities, and agricultural application. The effects of some factors on soil HMs showed a monotonic linear trend, but some have apparent threshold effects. The direction of influence on soil HMs will shift when pH and phosphate fertilizer reach a specific value. The addition of enterprises in the area would rarely have an impact on the HMs pollution once it reached around 2 per km2 because of the industrial agglomeration. Soil HM concentrations were mainly from multi-pollutants and were governed by a combination of environmental factors. Our study provided managers and policymakers with site-specific and definite guidelines for preventing and controlling soil HM pollution.
Source Identification and Apportionment of Potential Toxic Elements in Soils in an Eastern Industrial City, China.

Abstract:The extensive pattern of economic growth has an inestimable negative impact on the ecological environment, which causes the soil pollution problem to become increasingly prominent. In order to improve the effectiveness and rationality of prevention and control of heavy metal pollution in regional soil, it is necessary to understand the current situation of pollution, identify pollution sources and clarify future pollution risks. In this paper, an industrially developed city in eastern China was taken as the study region. The positive matrix factorization model (PMF) model and Unmix model was applied to identify and apportion the pollution sources of soil potential toxic elements after evaluating the ecological risk of soil potential toxic elements. The PMF model identified six factors, including single source and composite source. The Unmix model also identified six sources, including sources of nature, industrial discharge and traffic emissions. The comparison between the two models showed that Hg and Ni pollution, as well as Cr enrichment in the study region, were related to the industrial discharge from enterprises and factories. Cd pollution was related to traffic emission sources. Cu and Zn pollution were related to the multiple sources mixed with soil parent material, traffic emissions and industrial discharge from electronic enterprises. Pb pollution was related to natural sources (e.g., soil pH) but also to industrial sources (e.g., industrial wastes discharge). Enrichment was related to soil parent material and agricultural inputs. Our study also implies that soil heavy metal pollution or enrichment in the study region was mainly from anthropogenic sources and supplemented by natural sources.

Abstract:Petrochemical industry is a key industry of soil pollution, which presents great effects on human health and the ecological environment. It is of great significance to achieve rapid, economic and efficient health risk identification for petrochemical industry in China. In this work, an efficient method was developed based on extreme gradient boosting (XGBoost) algorithm for human health risk identification, which is different from the traditional health risk assessment with complicated procedures. In this methodology, an index system of 13 indicators was established from the perspective of "sources - pathways - receptors" for risk identification. The 10-fold cross validation was used to assess the generalization performance, and the accuracy, precision and recall were employed to evaluate the performance of the algorithms. Wilcoxon signed-rank test was conducted to analyze the differences between XGBoost and other models for statistical support. The results showed that XGBoost significantly presented a better performance for health risk identification over multilayer perceptron neural network with error backpropagation training (BPNN), support vector machine (SVM), gradient boosting decision tree (GBDT) and light gradient boosting machine (LightGBM), with an accuracy of 0.783. The most important features contributing to the risk identification were determined with the sequence of site location (in the industrial zone or not), site planning and production period. Great attention should be given to the petrochemical sites that are not located in the industrial zone with long production period and sensitive receptors in the health risk identification. This method has important reference significance for relevant departments to carry out soil contamination screening and health risk assessment of petrochemical sites.

Abstract:Heavy metal pollution in soil is threatening the ecological environment and human health. However, field measurement of heavy metal content in soil entails significant costs. Therefore, this study explores the estimation method of soil heavy metals based on remote sensing images and machine learning. To accurately estimate the heavy metal content, we propose a hybrid artificial intelligence model integrating least absolute shrinkage and selection operator (LASSO), genetic algorithm (GA) and error back propagation neural network (BPNN), namely the LASSO-GA-BPNN model. Meanwhile, this study compares the accuracy of the LASSO-GA-BPNN model, SVR (Support Vector Regression), RF (Random Forest) and spatial interpolation methods with Huanghua city as an example. Furthermore, the study uses the LASSO-GA-BPNN model to estimate the content of eight heavy metals (including Ni, Pb, Cr, Hg, Cd, As, Cu, and Zn) in Huanghua and visualize the results in high resolution. In addition, we calculate the Nemerow index based on the estimation results. The results denote that, the simultaneous optimization of BPNN by LASSO and GA can greatly improve the estimation accuracy and generalization ability. The LASSO-GA-BPNN model is a more accurate model for the estimate heavy metal content in soil compared to SVR, RF and spatial interpolation. Moreover, the comprehensive pollution level in Huanghua is mainly low pollution. The overall spatial distribution law of each heavy metal content is very similar, and the local spatial distribution of each heavy metal is different. The results are of great significance for soil pollution estimation.

Abstract:This study proposes a method for the rapid identification of elements in soil heavy metal pollution using spectral indices. Set up a simulation experiment of planting crops in soil polluted by multi-gradient Cu and Pb. The obtained polluted soil spectral data was initially pre-processed to obtain the original spectrum (OR), the continuum removed spectrum (CR), and the first-order differential spectrum (FOD). Then the preliminary model of soil heavy metal pollution index (SHMPI) was constructed. Using the correlation optimal algorithm, the maximum median distance algorithm, and the maximum average distance algorithm to select the optimal bands corresponding to the OR, CR, and FOD. The optimal bands selected by each algorithm were substituted into the SHMPI. Each algorithm obtains three indices, and two of them were selected as the x-axis and y-axis to form a two-dimensional pollution identification plane. Nine two-dimensional planes can be obtained by three algorithms and three combinations of OR, CR, and FOD. Support vector machine classifier was used to classify the Cu and Pb polluted samples in the planes, and nine classification models to distinguish Cu and Pb pollution in soil were constructed. The results show that using the correlation optimal algorithm to extract the optimal bands, and using OR and CR to construct SHMPI, the accuracy of the classification line model of Cu and Pb pollution obtained was 93% in the training group and 86% in the validation group. This method can stably and effectively identify the types of heavy metal pollution in soil, and can also effectively identify whether the soil is polluted by heavy metals, which is expected to guide the rapid and non-destructive identification of heavy metal pollution in polluted areas, and provide new ideas for the identification of other types of heavy metals in soil.

Abstract:Source apportionment can be an effective tool in mitigating soil pollution but its efficacy is often limited by a lack of information on the factors that influence the accumulation of pollutants at a site. In response to this limitation and focusing on a suite of heavy metals identified as priorities for pollution control, the study established a comprehensive pollution control framework using factor identification coupled with spatial agglomeration for agricultural soils in an industrialized part of Zhejiang Province, China. In addition to elucidating the key role of industrial and traffic activities on heavy metal accumulation through implementing a receptor model, specific influencing factors were identified using a random forest model. The distance from the soil sample location to the nearest likely industrial source was the most important factor in determining cadmium and copper concentrations, while distance to the nearest road was more important for lead and zinc pollution. Soil parent materials, pH, organic matter, and clay particle size were the key factors influencing accumulation of arsenic, chromium, and nickel. Spatial auto-correlation between levels of soil metal pollution and industrial agglomeration can enable a more targeted approach to pollution control measures. Overall, the approach and results provide a basis for improved accuracy in source apportionment, and thus improved soil pollution control, at the regional scale.

Abstract:Soil microplastic (MP) pollution has recently become increasingly aggravated, with severe consequences being generated. Understanding the spatial distribution characteristics of soil MPs is an important prerequisite for protecting and controlling soil pollution. However, determining the spatial distribution of soil MPs through a large number of soil field sampling and laboratory test analyses is unrealistic. In this study, we compared the accuracy and applicability of different machine learning models for predicting the spatial distribution of soil MPs. The support vector machine regression model with radial basis function (RBF) as kernel function (SVR-RBF) has a high prediction accuracy (R2 = 0.8934). Among the six ensemble models, random forest (R2 = 0.9007) could better explain the significance of source and sink factors affecting the occurrence of soil MPs. Soil texture, population density, and MPs point of interest (MPs-POI) were the main source-sink factors affecting the occurrence of soil MPs. Furthermore, the accumulation of MPs in soil was significantly affected by human activity. The spatial distribution map of soil MP pollution in the study area was drawn based on the bivariate local Moran's I model of soil MP pollution and the normalized difference vegetation index (NDVI) variation trend. A total of 48.74 km2 of soil was in an area of serious MP pollution, mainly concentrated in urban soil. This study provides a hybrid framework that includes spatial distribution prediction of MPs, source-sink analysis, and pollution risk area identification, providing scientific and systematic methods and techniques for pollution management in other soil environments.

Abstract:RecQ helicases play an essential role in maintaining genetic integrity in all organisms from Escherichia coli to humans. Defects to these enzymes are responsible for three distinct human diseases: Werner syndrome, Bloom syndrome and Rothmund-Thomson syndrome. All three diseases are characterized by a predisposition to cancer due to increased genomic instability. Previous studies on the effects of non-covalent DNA modifications on the catalytic activity of purified Werner and Bloom DNA helicases have shown that both enzymes have similar sensitivity profiles to these DNA-binding agents and are most strongly inhibited by the minor groove binder distamycin A. In this study, we show that the sensitivity profiles of E. coli RecQ to a number of DNA-binding ligands are different to those observed for WRN and Bloom helicases. These observations may give insights into the differences in molecular mechanisms underlying efficient motor function of RecQ helicases.

Abstract:Monitoring the spatial distribution and sources of heavy metals (HM) in soil is essential for avoiding health risks and achieving sustainable soil utilization. Multiple geospatial data, including remote sensing, climate, soil and topography data, were used to extract environmental covariates. Additionally, the spatial scene was employed as the alternative data of land use/land cover to describe the urban functions and human activity intensity in more detail. After converting to a uniform resolution of 30 m, these environmental covariates were adopted to characterize several common HM in soil, including copper (Cu), chromium (Cr), lead (Pb), nickel (Ni), and zinc (Zn). The RReliefF algorithm was used to identify several important variables. The quantification models of HM were established using back-propagation neural network (BPNN) and deep neural network (DNN). Besides, the impact of distance from the spatial scenes on HM were analyzed. The result demonstrated that the spatial scene is a key environmental covariate in estimating HM in soil. Compared with BPNN, the DNN model provided better accuracy (R 2 = 0.67–0.75) for estimation of five HM elements. Therefore, the DNN model was used to map HM concentrations at a grid scale of 30 m. The spatial scenes with the highest risk of HM pollution are industrial areas, residential areas, road, and commercial areas, and the concentration of HM is negatively correlated with the distance from these spatial scenes. The effective impact distances of industrial and residential areas are about 2000 m, and the effective impact distances of road and commercial areas are 500 m.

Abstract:From the perspective of the mechanism of soil pollution, it is difficult to explain the process of predicting the spatial distributions of soil heavy metal pollution using traditional geostatistical methods at a regional scale. Furthermore, few methods are available to proactively identify potential risk areas for preventing soil contamination. In this study, we selected 13 environmental factors related to the accumulation of soil heavy metals based on the source-sink theory. Then, the fuzzy k-means method in combination with the random forest (RF) method was used to classify potential risk areas. The concentrations and spatial distributions of the heavy metals were well predicted by RF, and the average values of the root mean square error of the prediction and R2 were 4.84 mg kg−1 and 0.57, respectively. The results indicated that the soil pH, fine particulate matter, and proximity to polluting enterprises significantly influenced the heavy metal pollution in soils, and the environmental variables varied significantly across the identified subregions. This study provides a theoretical basis for the sustainable management and control of soil pollution at the regional scale.
