Abstract:Video object detection (VOD) focuses on detecting objects for each frame in a video, which is a challenging task due to appearance deterioration in certain video frames. Recent works usually distill crucial information from multiple support frames to improve the reference features, but they only perform at frame level or proposal level that cannot integrate spatial-temporal features sufficiently. To deal with this challenge, we treat VOD as a spatial-temporal hierarchical features interacting process and introduce a Multi-level Spatial-Temporal (MST) feature aggregation framework to fully exploit frame-level, proposal-level, and instance-level information in a unified framework. Specifically, MST first measures context similarity in pixel space to enhance all frame-level features rather than only update reference features. The proposal-level feature aggregation then models object relation to augment reference object proposals. Furthermore, to filter out irrelevant information from other classes and backgrounds, we introduce an instance ID constraint to boost instance-level features by leveraging support object proposal features that belong to the same object. Besides, we propose a Deformable Feature Alignment (DAlign) module before MST to achieve a more accurate pixel-level spatial alignment for better feature aggregation. Extensive experiments are conducted on ImageNet VID and UAVDT datasets that demonstrate the superiority of our method over state-of-the-art (SOTA) methods. Our method achieves 83.3% and 62.1% with ResNet-101 on two datasets, outperforming SOTA MEGA by 0.4% and 2.7%.

Abstract:Detecting objects in surveillance videos is an important problem due to its wide applications in traffic control and public security. Existing methods tend to face performance degradation because of false positive or misalignment problems. We propose a novel framework, namely, Foreground Gating and Background Refining Network (FG-BR Net), for surveillance object detection (SOD). To reduce false positives in background regions, which is a critical problem in SOD, we introduce a new module that first subtracts the background of a video sequence and then generates high-quality region proposals. Unlike previous background subtraction methods that may wrongly remove the static foreground objects in a frame, a feedback connection from detection results to background subtraction process is proposed in our model to distill both static and moving objects in surveillance videos. Furthermore, we introduce another module, namely, the background refining stage, to refine the detection results with more accurate localizations. Pairwise non-local operations are adopted to cope with the misalignments between the features of original and background frames. Extensive experiments on real-world traffic surveillance benchmarks demonstrate the competitive performance of the proposed FG-BR Net. In particular, FG-BR Net ranks on the top among all the methods on hard and sunny subsets of the UA-DETRAC detection dataset, without any bells and whistles.
Relation Distillation Networks For Video Object Detection

Abstract:It has been well recognized that modeling object-toobject relations would be helpful for object detection. Nevertheless, the problem is not trivial especially when exploring the interactions between objects to boost video object detectors. The difficulty originates from the aspect that reliable object relations in a video should depend on not only the objects in the present frame but also all the supportive objects extracted over a long range span of the video. In this paper, we introduce a new design to capture the interactions across the objects in spatio-temporal context. Specifically, we present Relation Distillation Networks (RDN) - a new architecture that novelly aggregates and propagates object relation to augment object features for detection. Technically, object proposals are first generated via Region Proposal Networks (RPN). RDN then, on one hand, models object relation via multi-stage reasoning, and on the other, progressively distills relation through refining supportive object proposals with high objectness scores in a cascaded manner. The learnt relation verifies the efficacy on both improving object detection in each frame and box linking across frames. Extensive experiments are conducted on ImageNet VID dataset, and superior results are reported when comparing to state-of-the-art methods. More remarkably, our RDN achieves 81.8% and 83.2% mAP with ResNet-101 and ResNeXt-101, respectively. When further equipped with linking and rescoring, we obtain to-date the best reported mAP of 83.8% and 84.7%.
Depth Cue Enhancement and Guidance Network for RGB-D Salient Object Detection

Abstract:Depth maps have been proven profitable to provide supplements for salient object detection in recent years. However, most RGB-D salient object detection approaches ignore that there are usually low-quality depth maps, which will inevitably result in unsatisfactory results. In this paper, we propose a depth cue enhancement and guidance network (DEGNet) for RGB-D salient object detection by exploring the depth quality enhancement and utilizing the depth cue guidance to generate predictions with highlighted objects and suppressed backgrounds. Specifically, a depth cue enhancement module is designed to generate high-quality depth maps by enhancing the contrast between the foreground and the background. Then considering the different characteristics of unimodal RGB and depth features, we use different feature enhancement strategies to strengthen the representation capability of side-output unimodal features. Moreover, we propose a depth-guided feature fusion module to excavate depth cues provided by the depth stream to guide the fusion of multi-modal features by fully making use of different modal properties, thus generating discriminative cross-modal features. Besides, we aggregate cross-modal features at different levels to obtain the final prediction by adopting a pyramid feature shrinking structure. Experimental results on six benchmark datasets demonstrate that the proposed network DEGNet outperforms 17 state-of-the-art methods.
Spatial-Temporal Feature Aggregation Network for Video Object Detection

Abstract:Video object detection is a challenging problem in computer vision. In this paper, we propose a novel spatial-temporal feature aggregation network to deal with this issue. Specifically, we present a novel instance-level feature aggregation module as complementary to traditional pixel-level feature aggregation, in which we build a new movement estimation module to learn instance movements across frames. Then the Graph Convolutional Networks (GCNs) is applied to obtain temporal relation among instances over frames to implement instance-level feature aggregation. At last, we combine pixel-level and instance-level features by learnable soft weights to make use of their complementary information. Our framework is simple to implement and enables end-to-end training, which achieves state-of-art performance on the ImageNet VID dataset by extensive experiments.

Abstract:Although it is well believed for years that modeling relations between objects would help object recognition, there has not been evidence that the idea is working in the deep learning era. All state-of-the-art object detection systems still rely on recognizing object instances individually, without exploiting their relations during learning. This work proposes an object relation module. It processes a set of objects simultaneously through interaction between their appearance feature and geometry, thus allowing modeling of their relations. It is lightweight and in-place. It does not require additional supervision and is easy to embed in existing networks. It is shown effective on improving object recognition and duplicate removal steps in the modern object detection pipeline. It verifies the efficacy of modeling object relations in CNN based detection. It gives rise to the first fully end-to-end object detector.

Abstract:RGB-D salient object detection (RGB-D SOD) has currently attracted much attention for its prospect of broad application. On the basis of the "encoder-decoder" paradigm of the fully convolutional network (FCN), many FCN-based strategies have emerged and achieved huge progress, but underestimated the potential of level-specific characteristics of multi-modal features. In this paper, we propose the adaptive guided fusion network (AGFNet) to further mine the potential information between the depth image and the RGB image, and design an adaptive fusion and coarse-to-fine decoding strategy to achieve high-precision detection of salient objects. Specifically, we first use a two-stream encoder to extract the multi-level features of the RGB image and depth image but refrain from the previous practice of using depth features for each layer. Second, a simple but effective way named multi-modal selective fusion strategy is designed to fuse the multi-level features. Third, for enhancement of contextual information of each level adaptively, an adaptive cross fusion module (ACFM) fuses the features at all levels and outputs a coarse saliency map. Finally, a guided attention refinement module (GARM) utilizes the coarse saliency map to guide the final features from ACFM to realize the enhancement and obtain a refined saliency map. Our method is compared with other state-of-the-art RGB-SOD methods through extensive experiments, and the results demonstrate the superiority of our proposed AGFNet. Abstract:The authors report the case of a patient in whom a contralateral extradural hematoma developed immediately after craniotomy for a traumatic intracranial lesion. Contrary to other reported cases but one, intraoperative brain bulging was not observed in this case. The pathophysiology of this complication is discussed. Immediate postoperative CT scan in patients who do not improve as expected is recommended for the early detection of this complication.

Abstract:Salient object detection is a fundamental topic in computer vision. Previous methods based on RGB-D often suffer from the incompatibility of multi-modal feature fusion and the insufficiency of multi-scale feature aggregation. To tackle these two dilemmas, we propose a novel multi-modal and multi-scale refined network (M2RNet). Three essential components are presented in this network. The nested dual attention module (NDAM) explicitly exploits the combined features of RGB and depth flows. The adjacent interactive aggregation module (AIAM) gradually integrates the neighbor features of high, middle and low levels. The joint hybrid optimization loss (JHOL) makes the predictions have a prominent outline. Extensive experiments demonstrate that our method outperforms other state-of-the-art approaches.

Abstract:With the supplement of texture and geometry cues in depth maps, salient object detection (SOD) shifts from 2D to 3D, aiming to detect the most attractive object in a pair of color and depth images. Previous work primarily focused on regional integrity. Few methods are used to improve the edge quality of prediction results, resulting in a final prediction with a complete structure but blurred edges. Moreover, due to the complexity of real-life scenarios, the problem of effectively separating the salient object from complex background has become a hot potato. Aiming to address these issues, we propose a novel network, EGA-Net, to improve the edge quality and highlight the main features of the salient object. Specifically, in the EGA-Net, we propose a feature interaction (FI) module and an edge feature enhancement (EFE) module, respectively. Among them, the FI module is used to remove unimodal feature redundancy, capture multi-modal feature complementarity, and reduce the contamination of low-quality depth maps. The EFE is used to improve the edge quality of the final salient object prediction results. Furthermore, a Global Information Guide Integration (GIGI) module has been proposed to suppress the background noise and effectively highlight the salient objects' main features. It uses interleaving and fusion methods to automatically select and enhance the vital information in the original input features under the guidance of global features. We put the training of EGA-Net under the supervision of a new hybrid loss function that can simultaneously take global pixel point, foreground, and depth map quality into account. Quantitative and qualitative experiment results demonstrate that our method outperforms the 19 advanced methods on eight publicly available RGB-D salient object detection datasets with five evaluation metrics. Abstract:In this work, we introduce FARP-Net, an adaptive local-global feature aggregation and relation-aware proposal network for high-quality 3D object detection from pure point clouds. Our key insight is that learning adaptive local-global feature aggregation from an irregular yet sparse point cloud and generating superb proposals are both pivotal for detection. Technically, we propose a novel local-global feature aggregation layer (LGFAL) that fully exploits the complementary correlation between local features and global features, and fuses their strengths adaptively via an attention-based fusion module. Furthermore, we incorporate a lightweight feature affine module (LFAM) into LGFAL to map the local features into a normal distribution, thus acquiring fine-grained features of each local region in a weight-sharing manner. During object proposal generation, we propose a weighted relation-aware proposal module (WRPM) that uses an objectness-aware formalism to weigh the relation importance among object candidates for a clear and principal context, thereby facilitating the generation of high-quality proposals. The WRPM challenges the traditional practice of extracting contextual information among all object candidates, which is inefficient as object candidates are always noisy and redundant. Experimentally, FARP-Net delivers superior performance on two widely used benchmarks with fewer parameters, 64.0% mAP@0.25 on the SUN RGB-D dataset and 70.9% mAP@0.25 on the ScanNet V2 dataset. We further validate that the proposed LGFAL and WRPM can be integrated into both indoor and outdoor detectors to boost performance. The code is available at https://github.com/XT-1997/FARP-Net.

Graph Fusion Network for Multi-Oriented Object Detection

Abstract:In object detection, non-maximum suppression (NMS) methods are extensively adopted to remove horizontal duplicates of detected dense boxes for generating final object instances. However, due to the degraded quality of dense detection boxes and not explicit exploration of the context information, existing NMS methods via simple intersection-over-union (IoU) metrics tend to underperform on multi-oriented and long-size objects detection. Distinguishing with general NMS methods via duplicate removal, we propose a novel graph fusion network, named GFNet, for multi-oriented object detection. Our GFNet is extensible and adaptively fuse dense detection boxes to detect more accurate and holistic multi-oriented object instances. Specifically, we first adopt a locality-aware clustering algorithm to group dense detection boxes into different clusters. We will construct an instance sub-graph for the detection boxes belonging to one cluster. Then, we propose a graph-based fusion network via Graph Convolutional Network (GCN) to learn to reason and fuse the detection boxes for generating final instance boxes. Extensive experiments both on public available multi-oriented text datasets (including MSRA-TD500, ICDAR2015, ICDAR2017-MLT) and multi-oriented object datasets (DOTA) verify the effectiveness and robustness of our method against general NMS methods in multi-oriented object detection.

Video Relation Detection with Spatio-Temporal Graph

Abstract:What we perceive from visual content are not only collections of objects but the interactions between them. Visual relations, denoted by the triplet , could convey a wealth of information for visual understanding. Different from static images and because of the additional temporal channel, dynamic relations in videos are often correlated in both spatial and temporal dimensions, which make the relation detection in videos a more complex and challenging task. In this paper, we abstract videos into fully-connected spatial-temporal graphs. We pass message and conduct reasoning in these 3D graphs with a novel VidVRD model using graph convolution network. Our model can take advantage of spatial-temporal contextual cues to make better predictions on objects as well as their dynamic relationships. Furthermore, an online association method with a siamese network is proposed for accurate relation instances association. By combining our model (VRD-GCN) and the proposed association method, our framework for video relation detection achieves the best performance in the latest benchmarks. We validate our approach on benchmark ImageNet-VidVRD dataset. The experimental results show that our framework outperforms the state-of-the-art by a large margin and a series of ablation studies demonstrate our method's effectiveness.

Abstract:With the development of artificial intelligence technology, visual scene understanding has become a hot research topic. Online visual relation detection plays an important role in dynamic visual scene understanding. However, the complete modeling of dynamic relations and how to utilize a large amount of video content to infer visual relations are two difficult problems needed to be solved. Therefore, we propose Hierarchical Multi-Modal Fusion network for online video visual relation detection. We propose ASE-GCN to model dynamic scenes from different perspectives in order to fully capture visual relations in dynamic scenes. Meanwhile, we use trajectory features and natural language features as additional auxiliary features to describe the visual scene together with high-level visual features constructed by ASE-GCN. In order to make full use of these information to infer the visual relation, we design Hierarchical Fusion module before the relation predictor, which fuses the multi-role and multi-modal features using the methods based on attention and trilinear pooling. Comparative experiments on the ImageNet-VidVRD dataset demonstrate that our network outperforms other methods, while ablation studies verify the proposed modules are effective.

Abstract:We tackle the challenging problem of human-object interaction (HOI) detection. Existing methods either recognize the interaction of each human-object pair in isolation or perform joint inference based on complex appearance-based features. In this paper, we leverage an abstract spatial-semantic representation to describe each human-object pair and aggregate the contextual information of the scene via a dual relation graph (one human-centric and one object-centric). Our proposed dual relation graph effectively captures discriminative cues from the scene to resolve ambiguity from local predictions. Our model is conceptually simple and leads to favorable results compared to the state-of-the-art HOI detection algorithms on two large-scale benchmark datasets.
Modal-Adaptive Gated Recoding Network for RGB-D Salient Object Detection

Abstract:The multi-modal salient object detection model based on RGB-D information has better robustness in the real world. However, it remains nontrivial to better adaptively balance effective multi-modal information in the feature fusion phase. In this letter, we propose a novel gated recoding network (GRNet) to evaluate the information validity of the two modes, and balance their influence. Our framework is divided into three phases: perception phase, recoding mixing phase and feature integration phase. First, A perception encoder is adopted to extract multi-level single-modal features, which lays the foundation for multi-modal semantic comparative analysis. Then, a modal-adaptive gate unit (MGU) is proposed to suppress the invalid information and transfer the effective modal features to the recoding mixer and the hybrid branch decoder. The recoding mixer is responsible for recoding and mixing the balanced multi-modal information. Finally, the hybrid branch decoder completes the multi-level feature integration under the guidance of an optional edge guidance stream (OEGS). Experiments and analysis on eight popular benchmarks verify that our framework performs favorably against 9 state-of-art methods.

Depth-Guided Progressive Network for Object Detection

Abstract:Multi-scale object detection in natural scenes is still challenging. To enhance the multi-scale perception capability, some algorithms combine the lower-level and higher-level information via multi-scale feature fusion strategies. However, the inherent spatial properties among instances and relations between foreground and background are ignored. In addition, the human-defined "center-based" regression quality evaluation strategy, predicting a high-to-low score based on a linear relationship with the distance to the center of ground-truth box, is not robust to scale-variant objects. In this work, we propose a Depth-Guided Progressive Network (DGPNet) for multi-scale object detection. Specifically, besides the prediction of classification and localization, the depth is estimated and used to guide the image features in a weighted manner to obtain a better spatial representation. Therefore, depth estimation and 2D object detection are simultaneously learned via a unified network, where the depth features are merged as auxiliary information into the detection branch to enhance the discrimination among multi-scale objects. Moreover, to overcome the difficulty of empirically fitting the localization quality function, high-quality predicted boxes on scale-variant objects are more adaptively obtained by an IoU-aware progressive sampling strategy. We divide the sampling process into two stages, i.e., "statistical-aware" and "IoU-aware". The former selects thresholds for positive samples based on statistical characteristics of multi-scale instances, and the latter further selects high-quality samples by IoU on the basis of the former. Therefore, the final ranking scores better reflect the quality of localization. Experiments verify that our method outperforms state-of-the-art methods on the KINS and Cityscapes dataset.

Fianet: Video Object Detection Via Joint Feature-Level and Instance-Level Aggregation

Abstract:Video object detection task is challenging due to the nonrigid and rigid appearance deformations in videos. Most of the typical competitive methods are to enhance per-frame features through aggregating lots of previous and future frames. But feature-level aggregation isn’t robust to rigid deformations such as occlusion and rare postures. In this paper, we propose an online video object detection method with joint feature-level aggregation and instance-level aggregation network (FIANet). Besides feature-level aggregation, we design a spatial-temporal instance calibration module (STIC) to aggregate the instance as a whole, which can reduce the interference of local distorted and missed pixels. Joint featurelevel and instance-level aggregation can work collaboratively to overcome different deformations. Only using less previous frames, our method can achieve 81.6% mAP with relatively high speed on ImageNet VID, which is state-of-the-art compared with causal and non-causal methods.
HRYNet: A Highly Robust YOLO Network for Complex Road Traffic Object Detection

Abstract:Object detection is a crucial component of the perception system in autonomous driving. However, the road scene presents a highly intricate environment where the visibility and characteristics of traffic targets are susceptible to attenuation and loss due to various complex road scenarios such as lighting conditions, weather conditions, time of day, background elements, and traffic density. Nevertheless, the current object detection network must exhibit more learning capabilities when detecting such targets. This also exacerbates the loss of features during the feature extraction and fusion process, significantly compromising the network's detection performance on traffic targets. This paper presents a novel methodology by which to overcome the concerns above, namely HRYNet. Firstly, a dual fusion gradual pyramid structure (DFGPN) is introduced, which employs a two-stage gradient fusion strategy to enhance the generation of more comprehensive multi-scale high-level semantic information, strengthen the interconnection between non-adjacent feature layers, and reduce the information gap that exists between them. HRYNet introduces an anti-interference feature extraction module, the residual multi-head self-attention mechanism (RMA). RMA enhances the target information by implementing a characteristic channel weighting policy, thereby reducing background interference and improving the attention capability of the network. Finally, the detection performance of HRYNet was evaluated by utilizing three datasets: the horizontally collected dataset BDD1000K, the UAV high-altitude dataset Visdrone, and a custom dataset. Experimental results demonstrate that HRYNet achieves a higher mAP_0.5 compared with YOLOv8s on the three datasets, with increases of 10.8%, 16.7%, and 5.5%, respectively. To optimize HRYNet for mobile devices, this study presents Lightweight HRYNet (LHRYNet), which effectively reduces the number of model parameters by 2 million. The results demonstrate that LHRYNet outperforms YOLOv8s in terms of mAP_0.5, with improvements of 6.7%, 10.9%, and 2.5% observed on the three datasets, respectively.

Abstract:The human brain can effortlessly recognize and localize objects, whereas current 3D object detection methods based on LiDAR point clouds still report inferior performance for detecting occluded and distant objects: The point cloud appearance varies greatly due to occlusion, and has inherent variance in point densities along the distance to sensors. Therefore, designing feature representations robust to such point clouds is critical. Inspired by human associative recognition, we propose a novel 3D detection framework that associates intact features for objects via domain adaptation. We bridge the gap between the perceptual domain, where features are derived from real scenes with sub-optimal representations, and the conceptual domain, where features are extracted from augmented scenes that consist of non-occlusion objects with rich detailed information. A feasible method is investigated to construct conceptual scenes without external datasets. We further introduce an attention-based re-weighting module that adaptively strengthens the feature adaptation of more informative regions. The network's feature enhancement ability is exploited without introducing extra cost during inference, which is plug-and-play in various 3D detection frameworks. We achieve new state-of-the-art performance on the KITTI 3D detection benchmark in both accuracy and speed. Experiments on nuScenes and Waymo datasets also validate the versatility of our method.
