Abstract:Heart diseases are common diseases which affects the human health. The arrhythmias, which might not be critically life-threatening but still, need attention and therapy to avoid deterioration. There is no fast and accurate method to analyse ECG signal. In this paper a new approach is designed for heartbeat classification based on DWT and RBF neural network. Discrete Wavelet transform will be applied separately to each heartbeat to extract static features. In addition, RR interval information like QRS points is computed to provide dynamic features. These two different types of features are concatenated as feature vector and a Radial Basis Function Neural Network classifier is utilized for the classification of heartbeats into one of different classes. The work is done on the data from two ECG leads and both decisions are fused for the final classification decision. It will be validated on the baseline MIT/BIH arrhythmia database for accuracy and different performance parameter. The clinical results are compared for diagnosis. The result of the work gives an automatic heartbeat classification.

Abstract:Artificial intelligence (AI) aided cardiac arrhythmia (CA) classification has been an emerging research topic. Existing AI-based classification methods commonly analyze electrocardiogram (ECG) signals in lower dimensions, using one-dimensional (1D) temporal signals or two-dimensional (2D) images, which, however, may have limited capability in characterizing lead-wise spatiotemporal correlations, which are critical to the classification accuracy. In addition, existing methods mostly assume that the ECG data are linear temporal signals. This assumption may not accurately represent the nonlinear, nonstationary nature of the cardiac electrophysiological process. In this work, we have developed a three-dimensional (3D) recurrence plot (RP)-based deep learning algorithm to explore the nonlinear recurrent features of ECG and Vectorcardiography (VCG) signals, aiming to improve the arrhythmia classification performance. The 3D ECG/VCG images are generated from standard 12 lead ECG and 3 lead VCG signals for neural network training, validation, and testing. The superiority and effectiveness of the proposed method are validated by various experiments. Based on the PTB-XL dataset, the proposed method achieved an average F1 score of 0.9254 for the 3D ECG-based case and 0.9350 for the 3D VCG-based case. In contrast, recently published 1D and 2D ECG-based CA classification methods yielded lower average F1 scores of 0.843 and 0.9015, respectively. Thus, the improved performance and visual interpretability make the proposed 3D RP-based method appealing for practical CA classification.

Abstract:Sudden cardiac death remains a significant concern, emphasizing the critical need for intelligent diagnostic techniques in cardiac disease detection. Cardiologic Vascular Diseases (CVD) pose a significant global health challenge, often associated with unhealthy lifestyle habits. Electrocardiogram (ECG) monitoring plays a crucial role in assessing heart function, but its interpretation can be challenging due to signal complexity. This study proposes a novel approach utilizing fused Slantlet-Spatial features alongside Auto Regression (AR) coefficients to classify electrocardiogram (ECG) signals. Leveraging the Slantlet Transform (SLT) for its superior time localization capabilities and the simplicity of AR coefficients, this methodology aims to enhance the accuracy of cardiac illness classification. Nineteen distinct features were extracted from 300 ECG signals, each comprising 512 samples, enriching the classification scheme's efficacy. The fused feature extraction technique demonstrated success in improving overall accuracy. Employing Binary Particle Swarm Optimization (BPSO), irrelevant features were pruned, resulting in a refined feature vector of only 14 relevant features. This reduction in feature dimensionality significantly influenced the classification accuracy. Subsequently, the refined feature vector was introduced to the classification stage, employing four distinct classifiers: Support Vector Machine (SVM) with various kernel functions, K-Nearest Neighbors (K-NN), Naïve Bayes (NB), and Decision Tree (DT). Simulation results revealed the feasibility of achieving an average classification accuracy of 99.67% across ECG signal categories. Notably, the polynomial kernel function-SVM classifier, with only 2-fold cross-validation, yielded optimal performance. This study emphasizes the potential of fused Slantlet-Spatial and AR features in enhancing the accuracy of cardiac disease classification. Moreover, the efficacy of BPSO in feature selection and the superior performance of the SVM classifier highlight promising avenues for further research in intelligent cardiac diagnosis systems. The proposed approach outperforms existing methods and contributes to the early detection of cardiovascular abnormalities, potentially improving patient outcomes.

Abstract:In the article ECG signals both normal and arrhythmia are studied with different nonlinear methods including chaotic attractor, RPS, correlation dimension, etc, to revealing the connection between ECG signals and heart rhythm conditions from nonlinear view. The results indicate that when heart rhythm state changes, the projection of ECG signals attractors in RPS changes remarkably, which corresponds with clinic diagnosis. Relating to results from correlation dimension combined with SVD, some certain pattern can be discovered. Meanwhile, the nonlinear dynamic process of the changing heart rhythm state is discussed to have a new sight into some kind of heart rhythm from nonlinear theory, in contrast to the clinic physiological characters. The results can be reference for intelligent diagnosis of heart disease.

Abstract:The new design method of the automated classifying system for electrocardiograms recognition (ECG) of healthy and ill patients, based only on high-frequency components of ECG signal with the use of statistical images recognition is offered. Cardiograms of two groups of patients were studied: healthy and those who came through myocardial infarction. The first step of classification method is ECG wavelet decomposition to the 4th level and allocation of four high-frequency ECG components. The choice of the 4th decomposing level is explained by the fact that the first four high-frequency components represent high ECG frequencies from 30 to 350 Hz, and low-frequency component represents the undistorted smoothed ECG signal cleared of high-frequency oscillations. In case of more deep signal expansion the following high-frequency component has frequency spectrum to 30 Hz, and low frequency component is significantly distorted. For each of the first four components of wavelet decomposition there is a number of ECG numerical signs, including energy, entropy and frequency characteristics, 21 signs in total. During the second step reduction of the dimensionality of the feature space by using scatter matrix is made for two chosen ECG groups. It has turned out that the reduced feature space is one-dimensional. Histograms of values of this one-dimensional feature for groups of healthy and ill patients are constructed. The third step is finding of the dividing constant which is able to distinguish both groups of ECG records. For testing 96 ECG records of patients with normal cardiograms and 120 ECG records of the patients who came through myocardial infarction are used. Only three features (3%) of 96 given features values of the first group are referred by the classifier to patients group and only 20 features (< 17%) of 120 given features values of the second patients group are referred by the classifier to ECG group of healthy patients. Considering that for each patient the system determines 12 features by 12 standard assignments, testing results show well classification accuracy.

Abstract:Classification and prediction of heart disease is a significant problem to realize medical treatment and life protection. In this paper, persistent homology is involved to analyze electrocardiograms and a novel heart disease classification method is proposed. Each electrocardiogram becomes a point cloud by sliding windows and fast Fourier transform embedding. The obtained point cloud reveals periodicity and stability characteristics of electrocardiograms. By persistent homology, three features including normalized persistent entropy, maximum life of time and maximum life of Betty number are extracted. These features show the structural differences between different types of electrocardiograms and display encouraging potentiality in classification of heart disease.

Abstract:Contextual cues are predictive and provide behaviorally relevant information; they are not the main objective of the current task but can make behavior more efficient. Using fMRI, we investigated the brain networks involved in representing contextual information and translating it into an attentional control signal. Human subjects performed a visual search task for a low-contrast target accompanied by a single non-target that was either perceptually similar or more salient (i.e., higher contrast). Shorter reaction times (RTs) and higher accuracy were found on salient trials, suggesting that the salient item was rapidly identified as a non-target and immediately acts as a spatial “anti-cue” to reorient attention to the target. The relative saliency of the non-target determined BOLD responses in the left temporoparietal junction (TPJ) and inferior frontal gyrus (IFG). IFG correlated with RT specifically on salient non-target trials. In contrast, bilateral dorsal frontoparietal regions [including the frontal eye fields (FEFs)] were correlated with RT in all conditions. Effective connectivity analyses using dynamic causal modeling found an excitatory pathway from TPJ to IFG to FEF, suggesting that this was the pathway by which the contextual cue was translated into an attentional control signal that facilitated behavior. Additionally, the connection from FEF to TPJ was negatively modulated during target-similar trials, consistent with the inhibition of TPJ by dorsal attentional control regions during top-down serial visual search. We conclude that left TPJ and IFG form a sensory-driven network that integrates contextual knowledge with ongoing sensory information to provide an attentional control signal to FEF.
Exploring a new frontier in cardiac diagnosis: ECG analysis enhanced by machine learning and parametric quartic spline modeling

Abstract:The heart's study holds paramount importance in human physiology, driving valuable research in cardiovascular health. However, assessing Electrocardiogram (ECG) analysis techniques poses challenges due to noise and artifacts in authentic recordings. The advent of machine learning systems for automated diagnosis has heightened the demand for extensive data, yet accessing medical data is hindered by privacy concerns. Consequently, generating artificial ECG signals faithful to real ones is a formidable task in biomedical signal processing. This paper introduces a method for ECG signal modeling using parametric quartic splines and generating a new dataset based on the modeled signals. Additionally, it explores ECG classification using three machine learning techniques facilitated by Orange software, addressing both normal and abnormal sinus rhythms. The classification enables early detection and prediction of heart-related ailments, facilitating timely clinical interventions and improving patient outcomes. The assessment of synthetic signal quality is conducted through power spectrum analysis and cross-correlation analysis, power spectrum analysis of both real and synthetic ECG waves provides a quantitative assessment of their frequency content, aiding in the validation and evaluation of synthetic ECG signal generation techniques. Cross-correlation analysis revealing a robust correlation coefficient of 0.974 and precise alignment with a negligible time lag of 0.000 s between the synthetic and real ECG signals. Overall, the adoption of quartic spline interpolation in ECG modeling enhances the precision, smoothness, and fidelity of signal representation, thereby improving the effectiveness of diagnostic and analytical tasks in cardiology. Three prominent machine learning algorithms, namely Decision Tree, Logistic Regression, and Gradient Boosting, effectively classify the modeled ECG signals with classification accuracies of 0.98620, 0.98965, and 0.99137, respectively. Notably, all models exhibit robust performance, characterized by high AUC values and classification accuracy. While Gradient Boosting and Logistic Regression demonstrate marginally superior performance compared to the Decision Tree model across most metrics, all models showcase commendable efficacy in ECG signal classification. The study underscores the significance of accurate ECG modeling in health sciences and biomedical technology, offering enhanced accuracy and flexibility for improved cardiovascular health understanding and diagnostic tools.

Abstract:With heart health issues attracting much attention, wearable electrocardiogram (ECG) monitoring devices show a broad market prospect. This paper develops a generic ECG pre-processing algorithm and proposes a method for the single-lead ECG classification problem based on model stacking. Features such as RR-intervals, power spectrum, and higher-order statistics are computed and grouped into three classes. The support vector machine (SVM) classifier is trained separately based on each class of features, and subsequently, a fourth SVM classifier is trained on the prediction results of the three SVM classifiers at the first layer. To obtain more realistic results and better comparisons with previous studies, the algorithm follows the ANSI/AAMI EC57:2012 standard and is tested on a real ECG database. The experimental results show that the algorithm in this paper better overcomes the impact of the data imbalance problem and obtains good results.

Abstract:Early detection of arrhythmia and effective treatment can prevent deaths caused by cardiovascular disease (CVD). In clinical practice, the diagnosis is made by checking the electrocardiogram (ECG) beat-by-beat, but this is usually time-consuming and laborious. In the paper, we propose an automatic ECG classification method based on Continuous Wavelet Transform (CWT) and Convolutional Neural Network (CNN). CWT is used to decompose ECG signals to obtain different time-frequency components, and CNN is used to extract features from the 2D-scalogram composed of the above time-frequency components. Considering the surrounding R peak interval (also called RR interval) is also useful for the diagnosis of arrhythmia, four RR interval features are extracted and combined with the CNN features to input into a fully connected layer for ECG classification. By testing in the MIT-BIH arrhythmia database, our method achieves an overall performance of 70.75%, 67.47%, 68.76%, and 98.74% for positive predictive value, sensitivity, F1-score, and accuracy, respectively. Compared with existing methods, the overall F1-score of our method is increased by 4.75~16.85%. Because our method is simple and highly accurate, it can potentially be used as a clinical auxiliary diagnostic tool.

Identification of cardiovascular diseases through ECG classification using wavelet transformation

Abstract:Cardiovascular diseases are the leading cause of mortality globally, necessitating advancements in diagnostic techniques. This study explores the application of wavelet transformation for classifying electrocardiogram (ECG) signals to identify various cardiovascular conditions. Utilizing the MIT-BIH Arrhythmia Database, we employed both continuous and discrete wavelet transforms to decompose ECG signals into frequency sub-bands, from which we extracted eight statistical features per band. These features were then used to train and test various classifiers, including K-Nearest Neighbors and Support Vector Machines, among others. The classifiers demonstrated high efficacy, with some achieving an accuracy of up to 96% on test data, suggesting that wavelet-based feature extraction significantly enhances the prediction of cardiovascular abnormalities in ECG data. The findings advocate for further exploration of wavelet transforms in medical diagnostics to improve automation and accuracy in disease detection. Future work will focus on optimizing feature selection and classifier parameters to refine predictive performance further.

Abstract:Nowadays, automated analysis of the electrocardiogram (ECG) signal is a popular choice to facilitates easy and expert-independent detection of lethal cardiovascular diseases (CVDs). Although, a majority of the state-of-the-art algorithms are found to be lagging due to the use of complicated methodologies, limited dataset, high feature dimension, feature selection or intense classification techniques. In this research an original, easy-to-use ECG based methodology is proposed for completely automated identification of multiple types of critical CVDs. Primarily, after preprocessing the algorithm uses a simplified technique for exact detection of ECG fiducial points. Then, based on detected fiducial points, some well interpretable and prominent ECG time domain features are efficiently extracted and a binary feature matrix has been derived using those features from different leads. Finally, a distinctive score is evaluated from the binary feature matrix calculating the sum of weighted feature value and only by utilizing the score,discrimination between the various types of CVDs is highly detectable. Proficiency of the algorithm is widely evaluated on the 12-lead ECG signal data collected from Physikalisch-Technische-Bundesanstalt (PTB) and PTB-XL database. The algorithm presents promising outcome with average accuracy, sensitivity and specificity of 99.43%, 98.27% and 99.59%, respectively. Evidently, the algorithm is capable enough and efficient as well in comparison with other reported techniques till date. Moreover, the use of a unique score derived from the binary matrix ascertains the exact detection of multiple cardiac abnormalities and the superior classification accuracy makes the algorithm promising for personal computerized health monitoring applications.

Abstract:Cardiovascular is nowadays a common and threatening disease for humans. Computer-aided diagnostic (CAD) can diagnose cardiovascular by finding anomalies in an electrocardiogram (ECG). However, this conventional diagnostic approach is inefficient and needs extensive analysis and medical knowledge to diagnose accurately. Deep learning can help in the timely detection of anomalies. ECG being a multi-tone signal, CNN-based temporal features are not sufficient for classification. A classification can be improved by integrating multi-spectral information with temporal features. Furthermore, the one-dimension (1D) ECG signal needs complex preprocessing, including signal cleaning and RR peak detection, whereas deep CNN is more efficient for 2D signals. This paper proposes an automated CAD system for ECG classification using a 2D deep-convolution network (CNN). The proposed CNN uses multi-spectral information by integrating wavelet-based spectral features with CNN's temporal features. The 1D ECG is reshaped to a 2D image, and a wavelet-encoded 2D CNN is proposed to classify these 2D images into four classes. The proposed model is evaluated using MIT-BIH datasets containing two-channel ambulatory ECG signals. A comparative study of both 1D and 2D approaches using deep CNN is presented in the paper initially. Later, the proposed network is validated by evaluating various quantitative parameters using the MIT-BIH dataset, and a comparative analysis is shown. The proposed CNN outperformed other models achieving the highest accuracy of 99.52% and 95.64% F1 score. The study reveals that the proposed model avoids the complex preprocessing of the ECG signals of cleaning, RR point detection, and waveform cropping. Further integration of wavelet-based multi-spectral features in CNN has improved the classification accuracy.

Abstract:High frequency components of electrocardiogram are potentially useful for the diagnosis of heart diseases. But, until now, they have found only limited clinical applications because of the unsuccessful method of analysis. The Wigner-Ville Distribution (WVD) is a method jointly representing signals in the time and frequency domains. In this paper WVD was applied to the analysis of high frequency components of ECG with obtaining of some preliminary results. Abstract:Cardiovascular diseases have become more and more prominent in recent years, which have proven to be a major threat to people's health. Accurate detection of arrhythmia in patients has important implications for clinical treatment. The aim of this study was to propose a novel automatic classification method for arrhythmia in order to improve classification accuracy. The electrocardiogram (ECG) signal was subjected preprocessing for denoising purposes using a wavelet transform. Then, the local and global characteristics of the beat, which contained RR interval features according with the clinical diagnosis criterion, morphology features based on wavelet packet decomposition and statistical features along with kurtosis coefficient, skewness coefficient and variance are exploited and fused. Meanwhile, the dimensionality of wavelet packet coefficients were reduced via principal component analysis (PCA). Finally, these features were used as the input of the random forest classifier to train the model and were then compared with the support vector machine (SVM) and back propagation (BP) neural networks. Based on 100,647 beats from the MIT-BIH database, the proposed method achieved an average accuracy, specificity and sensitivity of 99.08%, 99.00% and 89.31%, respectively, using the intra-patient beats, and 92.31%, 89.98% and 37.47%, respectively, using the inter-patient beats. Moreover, two classification schemes, namely, inter-patient and intra-patient scheme, were validated. Compared with the other methods referred to in this paper, the performance of the novel method yielded better results.
Non-linear Analysis Based ECG Classification of Cardiovascular Disorders

Abstract:Multi-channel ECG-based cardiac disorders detection has an impact on cardiac care and treatment. Limitations of existing methods included variation in ECG waveforms due to the location of electrodes, high non-linearity in the signal, and amplitude measurement in millivolts. The present study reports a non-linear analysis-based methodology that utilizes Recurrence plot visualization. The patterned occurrence of well-defined structures, such as the QRS complex, can be exploited effectively using Recurrence plots. This Recurrence-based method is applied to the publicly available Physikalisch-Technische Bundesanstalt (PTB) dataset from PhysioNet database, where we studied four classes of different cardiac disorders (Myocardial infarction, Bundle branch blocks, Cardiomyopathy, and Dysrhythmia) and healthy controls, achieving an impressive classification accuracy of 100%. Additionally, t-SNE plot visualizations of the latent space embeddings derived from Recurrence plots and Recurrence Quantification Analysis features reveal a clear demarcation between the considered cardiac disorders and healthy individuals, demonstrating the potential of this approach.

Abstract:The human immunodeficiency virus type 1 (HIV-1) is extremely diverse. In assessing the utility of an HIV-1 vaccine, an important issue is the possibility of differential protection. We discuss statistical methods of inferring how the vaccine efficacy may vary with viral type from data that would be collected from a randomized, double-blind, placebo-controlled preventive vaccine efficacy trial. Detailed characterization of virus isolated from individuals infected during the trial will be available. We focus on the highly simplified case in which the viral characteristics are summarized by a single feature, which may be nominal, or a scalar quantity that represents distance between the isolate and the prototype virus or viruses used in the vaccine preparation. We consider discrete categorical and continuous response models for this quantity and identify models whose parameters can be interpreted as log ratios of strain-specific relative risks of infection in a prospective model for HIV-1 exposure and transmission. Methods of inference are described for the multinomial logistic regression (MLR) model for discrete categorical response, and a new semiparametric model which can be viewed as a continuous analog of the MLR model is introduced. The methods are illustrated by application to HIV-1 and hepatitis B vaccine trial data.
Two-stream Network for ECG Signal Classification

Abstract:Electrocardiogram (ECG), a technique for medical monitoring of cardiac activity, is an important method for identifying cardiovascular disease. However, analyzing the increasing quantity of ECG data consumes a lot of medical resources. This paper explores an effective algorithm for automatic classifications of multi-classes of heartbeat types based on ECG. Most neural network based methods target the individual heartbeats, ignoring the secrets embedded in the temporal sequence. And the ECG signal has temporal variation and unique individual characteristics, which means that the same type of ECG signal varies among patients under different physical conditions. A two-stream architecture is used in this paper and presents an enhanced version of ECG recognition based on this. The architecture achieves classification of holistic ECG signal and individual heartbeat and incorporates identified and temporal stream networks. Identified networks are used to extract features of individual heartbeats, while temporal networks aim to extract temporal correlations between heartbeats. Results on the MIT-BIH Arrhythmia Database demonstrate that the proposed algorithm performs an accuracy of 99.38\%. In addition, the proposed algorithm reaches an 88.07\% positive accuracy on massive data in real life, showing that the proposed algorithm can efficiently categorize different classes of heartbeat with high diagnostic performance.
