Abstract:Each type of soil has different optimal soil stabilisation additive content. To design the optimal soil stabilisation component, reliable and efficient models are required. The study proposes the Machine Learning (ML) model Support Vector Regression (SVR) to predict the Unconfined Compressive Strength (UCS) of stabilised soil. To be able to deliver optimal performance, five metaheuristic algorithms: Simulated Annealing (SA), Random Restart Hill Climbing (RRHC), Particle swarm optimisation (PSO), Hunger Games Search (HGS) and Slime Mould Algorithm (SMA) are integrated with the SVR model. To explore the effect of the number of inputs on the model's performance, the data was divided into two scenarios of input variable number. ML models are evaluated by K-Fold and numerical indicators R 2 , RMSE and MAE. The results show that in Scenario 1, the SVR-HGS model has a higher predictive performance than other predictive models. While in Scenario 2, the SVR-PSO model gives better performance than the remaining predictive models. SHapley Additive exPlanation (SHAP) and Partial Dependence Plots 2D (PDP) were used to gain insight into the effects of variables on UCS, and the effects of cement and lime on the variables. Obtaining variables that have an important influence on the variation of stabilised soil UCS, in which cement is considered the most significant variable. The detection of A-line value is a relatively important predictor of UCS. At a suitable A-line value, it is possible to reduce the content of chemical stabilising agents (cement, lime) while maintaining the UCS value at a relative threshold.

Abstract:The present work aims to propose a model for calculating unconfined compressive strength (UCS) of soil stabilized by geopolymer based on gene expression programming (GEP). The new model is compared with earlier models developed from artificial neural networks (ANN), multivariable regression analysis (MVR), multi-gene genetic programming (MGGP), and support vector machines (SVM) models. The results indicate that the GEP model is superior to MVR and MGGP models and quite comparable to ANN and SVM models. The study demonstrates the robustness of the GEP model through parametric analysis. Additionally, this model is simpler and easier to use in practice.

Abstract:Unconfined compressive strength (UCS) can be used to assess the applicability of geopolymer binders as ecologically friendly materials for geotechnical projects. Furthermore, soft computing technologies are necessary since experimental research is often challenging, expensive, and time-consuming. This article discusses the feasibility and the performance required to predict UCS using a Random Forest (RF) algorithm. The alkali activator studied was sodium hydroxide solution, and the considered geopolymer source material was ground-granulated blast-furnace slag and fly ash. A database with 283 clayey soil samples stabilized with geopolymer was considered to determine the UCS. The database was split into two sections for the development of the RF model: the training data set (80%) and the testing data set (20%). Several measures, including coefficient of determination (R), mean absolute error (MAE), and root mean square error (RMSE), were used to assess the effectiveness of the RF model. The statistical findings of this study demonstrated that the RF is a reliable model for predicting the UCS value of geopolymer-stabilized clayey soil. Furthermore, based on the obtained values of RMSE = 0.9815 and R2 = 0.9757 for the testing set, respectively, the RF approach showed to provide excellent results for predicting unknown data within the ranges of examined parameters. Finally, the SHapley Additive exPlanations (SHAP) analysis was implemented to identify the most influential inputs and to quantify their behavior of input variables on the UCS.

Abstract:The present research employs new boosting-based ensemble machine learning models i.e., gradient boosting (GB) and adaptive boosting (AdaBoost) to predict the unconfined compressive strength (UCS) of geopolymer stabilized clayey soil. The GB and AdaBoost models were developed and validated using 270 clayey soil samples stabilized with geopolymer, with ground-granulated blast-furnace slag and fly ash as source materials and sodium hydroxide solution as alkali activator. The database was randomly divided into training (80%) and testing (20%) sets for model development and validation. Several performance metrics, including coefficient of determination (R 2 ), mean absolute error (MAE), root mean square error (RMSE), and mean squared error (MSE), were utilized to assess the accuracy and reliability of the developed models. The statistical results of this research showed that the GB and AdaBoost are reliable models based on the obtained values of R 2 (= 0.980, 0.975), MAE (= 0.585, 0.655), RMSE (= 0.969, 1.088), and MSE (= 0.940, 1.185) for the testing dataset, respectively compared to the widely used artificial neural network, random forest, extreme gradient boosting, multivariable regression, and multi-gen genetic programming based models. Furthermore, the sensitivity analysis result shows that ground-granulated blast-furnace slag content was the key parameter affecting the UCS.

Abstract:It has been imperative to study and stabilize cohesive soils for use in the construction of pavement subgrade and compacted landfill liners considering their unconfined compressive strength (UCS). As long as natural cohesive soil falls below 200 kN/m2 in strength, there is a structural necessity to improve its mechanical property to be suitable for the intended structural purposes. Subgrades and landfills are important environmental geotechnics structures needing the attention of engineering services due to their role in protecting the environment from associated hazards. In this research project, a comparative study and suitability assessment of the best analysis has been conducted on the behavior of the unconfined compressive strength (UCS) of cohesive soil reconstituted with cement and lime and mechanically stabilized at optimal compaction using multiple ensemble-based machine learning classification and symbolic regression techniques. The ensemble-based ML classification techniques are the gradient boosting (GB), CN2, naïve bayes (NB), support vector machine (SVM), stochastic gradient descent (SGD), k-nearest neighbor (K-NN), decision tree (Tree) and random forest (RF) and the artificial neural network (ANN) and response surface methodology (RSM) to estimate the (UCS, MPa) of cohesive soil stabilized with cement and lime. The considered inputs were cement (C), lime (Li), liquid limit (LL), plasticity index (PI), optimum moisture content (OMC), and maximum dry density (MDD). A total of 190 mix entries were collected from experimental exercises and partitioned into 74-26% train-test dataset. At the end of the model exercises, it was found that both GB and K-NN models showed the same excellent accuracy of 95%, while CN2, SVM, and Tree models shared the same level of accuracy of about 90%. RF and SGD models showed fair accuracy level of about 65-80% and finally (NB) badly producing an unacceptable low accuracy of 13%. The ANN and the RSM also showed closely matched accuracy to the SVM and the Tree. Both of correlation matrix and sensitivity analysis indicated that UCS is greatly affected by MDD, then the consistency limits and cement content, and lime content comes in the third place while the impact of (OMC) is almost neglected. This outcome can be applied in the field to obtain optimal compacted for a lime reconstituted soil considering the almost negligible impact of compactive moisture.

Abstract:Unconfined compressive strength (UCS) is a critical property for assessing the engineering performances of sustainable materials, such as cement–fly ash mortar (CFAM), in the design of construction engineering projects. The experimental determination of UCS is time-consuming and expensive. Therefore, the present study aims to model the UCS of CFAM with boosting machine learning methods. First, an extensive database consisting of 395 experimental data points derived from the literature was developed. Then, three typical boosting machine learning models were employed to model the UCS based on the database, including gradient boosting regressor (GBR), light gradient boosting machine (LGBM), and Ada-Boost regressor (ABR). Additionally, the importance of different input parameters was quantitatively analyzed using the SHapley Additive exPlanations (SHAP) approach. Finally, the best boosting machine learning model's prediction accuracy was compared to ten other commonly used machine learning models. The results indicate that the GBR model outperformed the LGBM and ABR models in predicting the UCS of the CFAM. The GBR model demonstrated significant accuracy, with no significant difference between the measured and predicted UCS values. The SHAP interpretations revealed that the curing time (T) was the most critical feature influencing the UCS values. At the same time, the chemical composition of the fly ash, particularly Al2O3, was more influential than the fly-ash dosage (FAD) or water-to-binder ratio (W/B) in determining the UCS values. Overall, this study demonstrates that SHAP boosting machine learning technology can be a useful tool for modeling and predicting UCS values of CFAM with good accuracy. It could also be helpful for CFAM design by saving time and costs on experimental tests.

Abstract:The unconfined compressive strength (UCS) of alkali-activated slag (AAS)-based cemented paste backfill (CPB) is influenced by multiple design parameters. However, the experimental methods are limited to understanding the relationships between a single design parameter and the UCS, independently of each other. Although machine learning (ML) methods have proven efficient in understanding relationships between multiple parameters and the UCS of ordinary Portland cement (OPC)-based CPB, there is a lack of ML research on AAS-based CPB. In this study, two ensemble ML methods, comprising gradient boosting regression (GBR) and random forest (RF), were built on a dataset collected from literature alongside two other single ML methods, support vector regression (SVR) and artificial neural network (ANN). The results revealed that the ensemble learning methods outperformed the single learning methods in predicting the UCS of AAS-based CPB. Relative importance analysis based on the best-performing model (GBR) indicated that curing time and water-to-binder ratio were the most critical input parameters in the model. Finally, the GBR model with the highest accuracy was proposed for the UCS predictions of AAS-based CPB.

Data‐driven approach for investigating and predicting of compressive strength of fly ash–slag geopolymer concrete

Abstract:Fly ash–slag geopolymer concrete is an intangible material that does not use conventional Portland cement, thereby reducing CO2 emissions into the environment, and helping to increase sustainable development. However, compared with conventional concrete, the compressive strength of fly ash–slag geopolymer concrete is complexly dependent on many factors. Using the data‐driven approach for investigating and predicting fly ash–slag geopolymer concrete compressive strength is a suitable choice. This study introduces 11 easily accessible machine learning models in open‐source libraries of the Python programming language such as support vector machine, random forest (RF), gradient boosting (GB), AdaBoost, decision trees, light GB machine, extreme GB (XGB), K‐nearest neighbors, multivariable regression, Gaussian process regression, and CatBoost (CatB). Based on a dataset of 158 samples, 14 inputs, and 1 output variable compressive strength, the performance of 11 machine learning models was evaluated through 4 criteria including coefficient of determination, root mean square error, mean absolute error, and mean absolute percentage error combined with 10 repeats of 10‐fold cross‐validation. Four models have the best performance based on the above four criteria value in determining compressive strength for testing dataset sorted descending is CatB > XGB > RF > GB. Global Shapley (SHAP) value‐based CatB and XGB indicates three groups of factors with decreasing influence on compressive strength of geopolymer concrete: group I (slag, molarity, coarse aggregate, curing temperature, and alkaline activator/binder) > group II (Na2SiO3 content, NaOH content, fine aggregate, fly ash content), curing period > group III (extra water added, NaOH/Na2SiO3, superplasticizer content, rest period). Extra water added, NaOH/Na2SiO3, superplasticizer content, rest period have insignificant influence on the compressive strength value of geopolymer concrete. The greater the slag content in the slag–fly ash mixture, the greater the compressive strength of geopolymer concrete. The optimum molarity of NaOH concentration is about 14–16 M for designing the compressive strength of geopolymer concrete. SHAP values partial dependence plots (PDP) and PDP indicate that alkaline activator/binder optimal values exist to achieve high compressive strength. The compressive strength increases with curing temperature between 20 and 100°C. PDP values show that the tendency to increase compressive strength with increasing coarse aggregate content from about 750 to 1250 kg/m3.

Abstract:Machine learning (ML) techniques are often employed for the accurate prediction of the compressive strength of concrete. Despite higher accuracy, previous ML models failed to interpret the rationale behind predictions. Model interpretability is essential to appeal to the interest of domain experts. Therefore, overcoming research gaps identified, this research study proposes a way to predict the compressive strength of concrete using supervised ML algorithms (Decision tree, Extra tree, Adaptive boost (AdaBoost), Extreme gradient boost (XGBoost), Light gradient boosting method (LGBM), and Laplacian Kernel Ridge Regression (LKRR). Alternatively, SHapley Additive exPlainations (SHAP) – a novel black-box interpretation approach - was employed to elucidate the predictions. The comparison revealed that tree-based algorithms and LKRR provide acceptable accuracy for compressive strength predictions. Moreover, XGBoost and LKRR algorithms evinced superior performance (R = 0.98). According to SHAP interpretation, XGBoost predictions capture complex relationships among the constituents. On the other hand, SHAP provides unified measures on feature importance and the impact of a variable for a prediction. Interestingly, SHAP interpretations were in accordance with what is generally observed in the compressive behavior of concrete, thus validating the causality of ML predictions.

Abstract:This study proposed a procedure to optimize the mixture proportion of geopolymer using machine learning (ML) and multi-objective optimization (MOO) model, which enhances the compressive strength and minimizes the carbon emission and costs. The experiment was preliminary carried out to analyze the workability, compressive strength, microstructure, and pore characteristics of fly ash/slag-based geopolymer. The results showed that the higher replacement ratio of slag established positive effects on the hardening as well as porosity improvement due to the coexistence of C-S-H and NASH-type binders, especially for a ratio was no more than 60%. Considering the performance of geopolymers is often influenced by multiple factors such as material composition and curing conditions, which could not be solved by traditional methods. A database containing 836 samples was established to analyze the prediction performance of 7 ML models by using Bayesian optimization. The GPR model has good generalization ability, with R2 being 0.99 (0.99) on the testing set (training set). Furthermore, the reliability of the ML models was evaluated by the tests conducted in this paper. The feature importance analysis utilizing SHAP method indicates that Age, HM, and SS are key parameters influencing the compressive strength of geopolymer. The proposed MOO model can effectively evaluate the trade-offs between compressive strength, carbon emission, and costs, and all Pareto solutions for bi-objective and three-objective provided the optimal mixture schemes. On this basis, the design procedure proposed in this paper can give the scheme of geopolymer materials with different requirements (given mixture scheme and given design strength).
Modeling the influence of lime on the unconfined compressive strength of reconstituted graded soil using advanced machine learning approaches for subgrade and liner applications

Abstract:In the field of soil mechanics, especially in transportation and environmental geotechnics, the use of machine learning (ML) techniques has emerged as a powerful tool for predicting and understanding the compressive strength behavior of soils especially graded ones. This is to overcome the sophisticated equipment, laboratory space and cost needs utilized in multiple experiments on the treatment of soils for environmental geotechnics systems. This present study explores the application of machine learning (ML) techniques, namely Genetic Programming (GP), Artificial Neural Networks (ANN), Evolutionary Polynomial Regression (EPR), and the Response Surface Methodology in predicting the unconfined compressive strength (UCS) of soil-lime mixtures. This was for purposes of subgrade and landfill liner design and construction. By utilizing input variables such as Gravel, Sand, Silt, Clay, and Lime contents (G, S, M, C, L), the models forecasted the strength values after 7 and 28 days of curing. The accuracy of the developed models was compared, revealing that both ANN and EPR achieved a similar level of accuracy for UCS after 7 days, while the GP model performed slightly lower. The complexity of the formula required for predicting UCS after 28 days resulted in decreased accuracy. The ANN and EPR models achieved accuracies of 85% and 82%, with R 2 of 0.947 and 0.923, and average error of 0.15 and 0.18, respectively, while the GP model exhibited a lower accuracy of 66.0%. Conversely, the RSM produced models for the UCS with predicted R 2 of more than 98% and 99%, for the 7- and 28- day curing regimes, respectively. The RSM also produced adequate precision in modelling UCS of more than 14% against the standard 7%. All input factors were found to have almost equal importance, except for the lime content (L), which had an average influence. This shows the importance of soil gradation in the design and construction of subgrade and landfill liners. This research further demonstrates the potential of ML techniques for predicting the strength of lime reconstituted G-S-M-C graded soils and provides valuable insights for engineering applications in exact and sustainable subgrade and liner designs, construction and performance monitoring and rehabilitation of the constructed civil engineering infrastructure.

Mechanical Framework for Geopolymer Gels Construction: An Optimized LSTM Technique to Predict Compressive Strength of Fly Ash-Based Geopolymer Gels Concrete

Abstract:As an environmentally responsible alternative to conventional concrete, geopolymer concrete recycles previously used resources to prepare the cementitious component of the product. The challenging issue with employing geopolymer concrete in the building business is the absence of a standard mix design. According to the chemical composition of its components, this work proposes a thorough system or framework for estimating the compressive strength of fly ash-based geopolymer concrete (FAGC). It could be possible to construct a system for predicting the compressive strength of FAGC using soft computing methods, thereby avoiding the requirement for time-consuming and expensive experimental tests. A complete database of 162 compressive strength datasets was gathered from the research papers that were published between the years 2000 and 2020 and prepared to develop proposed models. To address the relationships between inputs and output variables, long short-term memory networks were deployed. Notably, the proposed model was examined using several soft computing methods. The modeling process incorporated 17 variables that affect the CSFAG, such as percentage of SiO2 (SiO2), percentage of Na2O (Na2O), percentage of CaO (CaO), percentage of Al2O3 (Al2O3), percentage of Fe2O3 (Fe2O3), fly ash (FA), coarse aggregate (CAgg), fine aggregate (FAgg), Sodium Hydroxide solution (SH), Sodium Silicate solution (SS), extra water (EW), superplasticizer (SP), SH concentration, percentage of SiO2 in SS, percentage of Na2O in SS, curing time, curing temperature that the proposed model was examined to several soft computing methods such as multi-layer perception neural network (MLPNN), Bayesian regularized neural network (BRNN), generalized feed-forward neural networks (GFNN), support vector regression (SVR), decision tree (DT), random forest (RF), and LSTM. Three main innovations of this study are using the LSTM model for predicting FAGC, optimizing the LSTM model by a new evolutionary algorithm called the marine predators algorithm (MPA), and considering the six new inputs in the modeling process, such as aggregate to total mass ratio, fine aggregate to total aggregate mass ratio, FASiO2:Al2O3 molar ratio, FA SiO2:Fe2O3 molar ratio, AA Na2O:SiO2 molar ratio, and the sum of SiO2, Al2O3, and Fe2O3 percent in FA. The performance capacity of LSTM-MPA was evaluated with other artificial intelligence models. The results indicate that the R2 and RMSE values for the proposed LSTM-MPA model were as follows: MLPNN (R2 = 0.896, RMSE = 3.745), BRNN (R2 = 0.931, RMSE = 2.785), GFFNN (R2 = 0.926, RMSE = 2.926), SVR-L (R2 = 0.921, RMSE = 3.017), SVR-P (R2 = 0.920, RMSE = 3.291), SVR-S (R2 = 0.934, RMSE = 2.823), SVR-RBF (R2 = 0.916, RMSE = 3.114), DT (R2 = 0.934, RMSE = 2.711), RF (R2 = 0.938, RMSE = 2.892), LSTM (R2 = 0.9725, RMSE = 1.7816), LSTM-MPA (R2 = 0.9940, RMSE = 0.8332), and LSTM-PSO (R2 = 0.9804, RMSE = 1.5221). Therefore, the proposed LSTM-MPA model can be employed as a reliable and accurate model for predicting CSFAG. Noteworthy, the results demonstrated the significance and influence of fly ash and sodium silicate solution chemical compositions on the compressive strength of FAGC. These variables could adequately present variations in the best mix designs discovered in earlier investigations. The suggested approach may also save time and money by accurately estimating the compressive strength of FAGC with low calcium content.

Abstract:The flyash-based geopolymer concrete has been extensively utilized to minimize carbon emissions for over 15 years. The compressive strength (CS), split tensile strength (STS), and flexural strength (FS) of concrete determine its mechanical characteristics. Laboratory strength testing and analytical methods is costly and time-consuming, which struggle to predict complicated concrete combination CS, STS, and FS. ML models accurately predict CS, STS, FS. To predict the CS, STS, and FS of GPC concrete, five ML techniques (LR, SVM, GPR, EL, and ANN) were adopted. Taylor diagrams and error graphs adopted to represents model performances. The GPR outperforms other models in CS predictions by having the lowest MAE, RMSE, MAPE, and R-values. GPR continues to outperform in STS predictions, with low MAE, RMSE, and MAPE, as well as high R-values. GPR outperforms FS predictions with low MAE, RMSE, MAPE, and high R-values. SVM is excellent since it has a low MAE and RMSE. SVM, GPR, and ANN optimisations keep them competitive. GPR consistently gets the lowest MAPE values across all three tests, indicating that it is a strong model contender. Abstract:This paper presents a novel application of machine learning models to clarify the intricate behaviors of expansive soils, focusing on the impact of sand content, saturation level, and dry density. Departing from conventional methods, this research utilizes a data-centric approach, employing a suite of sophisticated machine learning models to predict soil properties with remarkable precision. The inclusion of a 30% sand mixture is identified as a critical threshold for optimizing soil strength and stiffness, a finding that underscores the transformative potential of sand amendment in soil engineering. In a significant advancement, the study benchmarks the predictive power of several models including extreme gradient boosting (XGBoost), gradient boosting regression (GBR), random forest regression (RFR), decision tree regression (DTR), support vector regression (SVR), symbolic regression (SR), and artificial neural networks (ANNs and proposed ANN-GMDH). Symbolic regression equations have been developed to predict the elasticity modulus and unconfined compressive strength of the investigated expansive soil. Despite the complex behaviors of expansive soil, the trained models allow for optimally predicting the values of unconfined compressive parameters. As a result, this paper provides for the first time a reliable and simply applicable approach for estimating the unconfined compressive parameters of expansive soils. The proposed ANN-GMDH model emerges as the pre-eminent model, demonstrating exceptional accuracy with the best metrics. These results not only highlight the ANN’s superior performance but also mark this study as a groundbreaking endeavor in the application of machine learning to soil behavior prediction, setting a new benchmark in the field.

Using machine learning technique for designing reinforced lightweight soil

Abstract:Taking advantage of dredged sediments as lightweight materials is a useful solution to protect the environment and save natural materials in the field of construction. In which unconfined compression strength is an important criterion to determine the application in the construction project. It is difficult to find the optimal mixing ratio based on design standards or construction conditions because the unconfined compression strength (UCS) is affected by the mixing ratio of the materials and additives. In this study, the Machine Learning (ML) models consisting of Extreme Gradient Boosting (XGB) model and Linear regression models are investigated to design components for reinforced lightweight soil based on the influence of unconfined compression strength of the test sample which is water content, cement content, air foam content, waste fishing net. To evaluate the effectiveness of the proposed ML models, several evaluation criteria including Mean Absolute Error (MAE), Root Mean Square Error (RMSE) and coefficient of determination (R2) are proposed. The results show that the predictions of the XGB model have high accuracy with R2 = 0.9695, RMSE = 5.5849 kPa and MAE = 4.1583 kPa for the testing dataset. Sensitivity analysis evaluates the influence of input variables on UCS and the interaction between input variables to help design RLS components optimally.

Abstract:Supplementary cementitious materials (SCM) are key components of low-carbon cementitious materials. However, their effects, especially for the emerging high cement replacement ratio formulations, are sometimes very challenging to predict, leading to restrictions in most standards. Through advanced Machine Learning techniques, this study provides novel insights into the autogenous shrinkage properties of concrete containing various kinds of supplementary cementitious materials such as slag, fly ash, silica fume, calcined clay, and filler. Four machine learning models are optimized and their predictions are compared on a dedicated database, including ternary and quaternary cement blends. The Extreme Gradient Boosting (XGBoost) model exhibited the highest accuracy among these models. Interpretative tools such as SHAP analysis are then used to obtain novel information about the relative influence of the SCM on the autogenous shrinkage depending on their dosage. The model is finally compared to the recently modified versions of the B4 and the CEB analytical models to predict the autogenous shrinkage of unknown concrete formulations. The model showed significantly better predictions than the analytical models, and a web application is proposed, paving the way for precise and interpretable autogenous shrinkage predictions of cementitious materials incorporating SCM.

Abstract:In this study, a compressive strength prediction model for Magnesium Phosphate Cement containing solid waste materials (SW-MPC) was developed using machine learning (ML) techniques. Firstly, a database of SW-MPC compressive strength was established through the selection of solid waste materials based on their chemical compositions. Subsequently, various ML algorithms were employed to construct predictive models for SW-MPC compressive strength, and the predictive accuracy of these models was compared. Furthermore, Shapley Additive Explanations (SHAP) analysis was utilized to assess the impact of various parameters on SW-MPC compressive strength. The results revealed that the Extreme Gradient Boosting (XGB) model exhibited the highest predictive accuracy and generalization ability. Among numerous feature parameters, the curing age (Age) and phosphate type (Type_PO 4 ) were identified as the most critical factors influencing SW-MPC compressive strength. SW-MPC compressive strength exhibited a positive correlation with the Si content (Con_Si) and Al content (Con_Al) in the solid waste materials, while it generally displayed a negative correlation with Fe content (Con_Fe). The optimal Magnesium-to-Phosphorus ratio (M/P) for SW-MPC preparation ranged from 4 to 6. Furthermore, the influence of the dosage of solid waste materials (Per_sw) on the compressive strength of SW-MPC was complex, with the optimal content being around 10% and 35%. This complexity arose from the significant impact of the interactive effects between the content of different elements in solid waste materials and Per_sw on the compressive strength of SW-MPC.

Abstract:Geopolymer concrete (GPC) based on fly ash (FA) is being studied as a possible alternative solution with a lower environmental impact than Portland cement mixtures. However, the accuracy of the strength prediction still needs to be improved. This study was based on the investigation of various types of machine learning (ML) approaches to predict the compressive strength (C-S) of GPC. The support vector machine (SVM), multilayer perceptron (MLP), and XGBoost (XGB) techniques have been employed to check the difference between the experimental and predicted results of the C-S for the GPC. The coefficient of determination (R2) was used to measure how accurate the results were, which usually ranged from 0 to 1. The results show that the XGB was a more accurate model, indicating an R2 value of 0.98, as opposed to SVM (0.91) and MLP (0.88). The statistical checks and k-fold cross-validation (CV) also confirm the high precision level of the XGB model. The lesser values of the errors for the XGB approach, such as mean absolute error (MAE), mean square error (MSE), and root mean square error (RMSE), were noted as 1.49 MPa, 3.16 MPa, and 1.78 MPa, respectively. These lesser values of the errors also indicate the high precision of the XGB model. Moreover, the sensitivity analysis was also conducted to evaluate the parameter’s contribution towards the anticipation of C-S of GPC. The use of ML techniques for the prediction of material properties will not only reduce the effort of experimental work in the laboratory but also minimize the cast and time for the researchers.

Abstract:In this study, the properties of controlled low strength material (CLSM) made from waste soil were examined, utilizing 53 different mix proportions, and a dataset was subsequently constructed. Models, such as particle swarm optimization (PSO)-support vector regression (SVR), genetic algorithm (GA)-SVR, and grid search (GS)-SVR, were developed to predict both flowability and unconfined compressive strength (UCS). To assess the models' performance, comparisons between experimental and predicted values, residual distribution histograms, and evaluation criteria were conducted. Results revealed that all three models effectively predicted the flowability and UCS of CLSM made from waste soil. Predicted values closely aligned with experimental values in both training and testing sets. Notably, GA-SVR exhibited greater accuracy when compared to PSO-SVR and GS-SVR. Evaluation criteria, including correlation coefficient ( R 2 ), mean square error (MSE), root mean square error (RMSE), mean absolute error (MAE), and mean absolute percentage error (MAPE) for GA-SVR in assessing flowability were 0.948, 77.899, 8.826, 7.608, and 3.061 %, respectively. Correspondingly, for UCS, the values were 0.934, 0.032, 0.178, 0.115, and 8.956 %, respectively. Furthermore, the histogram depicting the residual distribution of the GA-SVR model closely resembled a normal distribution, characterized by a small mean and standard deviation. Extending the analysis to 45 compression strength data points obtained from public literature, the three models continued to demonstrate effective predictive capabilities, with the GA-SVR model outperforming the others. The evaluation criteria, including R 2 , MSE, RMSE, MAE, and MAPE in this context were 0.909, 0.011, 0.105, 0.085, and 15.502 %, respectively. Shapley additive explanation (SHAP) values highlighted water as the most crucial input variable in the flowability model. Additionally, water, superplasticizer (SP), and sand positively impacted flowability, whereas soil, fly ash (FA), and cement exerted negative effects. In the UCS model, curing age (CA) emerged as the most important input variable. CA, cement, FA, sand, and soil positively influenced UCS, while water and SP had negative effects. This study is of considerable importance in the accurate prediction and evaluation of CLSM engineering properties, as well as in optimizing mix proportions.

Abstract:Based on the heterogeneity of concrete constituents as well as variability in compressive strength over many magnitudes for various types of concrete, predictive methods for evaluating the compressive strength have now been given considerable attention. As a result, this research compares the performance of the Artificial Neural Network, ANN, in forecasting the compressive strength of geopolymer recycledconcrete (GPRC)based on selected pozzolans (Coal Fly Ash (CFA) and Rice Husk Ash (RHA)) at ages 7, 28, and 56 daysto the traditional Multiple Linear Regression, MLR. The compressive strength of GPRC-based CFAand RHA was determined using 65 concrete samples from eight different mixtures.The developed models were based on the experimental results, which used varying material quantities. The ANN and MLR models were built with eightinput variables: Ordinary Portland cement (OPC), RHA, CFA, Crushed granite (CG), Cupola Furnace Slag (CFS), Alkaline Solution (AS), Water-Binder Ratio (WB), and Concrete Age (CA), with compressive strength being the only predicted variable. Using MATLAB® code, approximately 75% and 25% of the input data were used for training and testing to develop an ANN model for predicting compressive strength, fcu.For ANN and MLR, the input data were trained and tested using the feedforward back-proportion and backward eliminationapproaches, respectively. Based on satisfactory performance in terms of means square error MSE, the most likely model architecture containing eight input layers, thirteen hidden layers, and one output layer neurons was chosen after several trials. According to the MLR results, only three input variables, CFA, CG, and CA, are statistically significant with p-values less than 0.05. R2= 0.9972, MSE = 0.4177, RMSE = 1.8201,for ANN and R2= 0.7410, MSE = 66.6308, RMSE = 290.4370, for MLR. The predicted results demonstrate the proposed model's dependability and computational forecasting capability. The findings of the study have the potential to help a wide range of construction industry in predicting the concrete properties and managing scarce resources.
