Abstract:Smart applications are appealing an accurate matching between users and items, in which recommendation technologies are applied widely. Since recommendation serve for two roles, namely users and items, accuracy is not the only focus, the diversification and fairness should also be paid more attention for improving recommendation performance. The tradeoff among the accuracy, diversification and fairness on recommendation is bringing a big challenge. This paper proposed a novelty recommendation model to ensure the recommendation performance, which introduces a multi-variate linear regression model to cooperate with the collaborative filtering method. This study utilizes an improved similarity metrics to discover the closeness between users and item categories under the help of the collaborative filtering methods, and exploits the micro attribute information of items by a multi-variate linear regression model to decide the final recommended items. The experimental results show that our proposed method can provide better recommendation accuracy, diversification and fairness than the recommendation based on pure collaborative filtering method.

Empirical Research on the Impact of Personalized Recommendation Diversity.

Abstract:Personalized recommendation has important implications in raising online shopping efficiency and increasing product sales. There has been wide interest in finding ways to provide more efficient personalized recommendations. Most existing studies focus on how to improve the accuracy of the recommendation algorithms, or are more concerned on ways to increase consumer satisfaction. Unlike these studies, our study focuses on the process of decision-making, using long tail theory as a basis, to reveal the mechanisms involved in consumers' adoption of recommendations. This paper analyzes the effect of personalized recommendations from two angles: product sales and ratings, and tries to point out differences in consumer preferences between mainstream products and niche products, high rating products and low rating products, search products and experience products. The study verifies that consumers demand diversity in the recommended content, and also provides suggestions on how to better plan and operate a personalized recommendation system.

Diversify or Not: Dynamic Diversification for Personalized Recommendation

Abstract:Diversity is believed to be an essential factor in improving user satisfaction in recommender systems, while how to take advantage of it has long been a problem worth exploring. Existing work either ignores the influence of diversity or overlooks users’ different diversity demands in recommendations. In this study, we analyze users’ behaviors on a real-world dataset collected from an e-commerce website and find that the demand for diversity changes among different users, even the same user’s demand varies among different shopping scenarios. There is also evidence that users’ behaviors are affected by the diversity of impressions, which has been often ignored by traditional session-based recommendation models. Then, we propose a Dynamic Diversification Recommendation Model (DDRM) with the integration of both click and impression diversities to better make use of diversity for recommendations. Extensive experimental results demonstrate that DDRM outperforms all baseline methods significantly. Further studies show our model can provide more precise and reasonable recommendations.

Abstract:Users of industrial recommender systems are normally suggesteda list of items at one time. Ideally, such list-wise recommendationshould provide diverse and relevant options to the users. However, in practice, list-wise recommendation is implemented as top-N recommendation. Top-N recommendation selects the first N items from candidates to display. The list is generated by a ranking function, which is learned from labeled data to optimize <a class="link-external link-http" href="http://accuracy.However" rel="external noopener nofollow">this http URL</a>, top-N recommendation may lead to suboptimal, as it focuses on accuracy of each individual item independently and overlooks mutual influence between items. Therefore, we propose a personalized re-ranking model for improving diversity of the recommendation list in real recommender systems. The proposed re-ranking model can be easily deployed as a follow-up component after any existing ranking function. The re-ranking model improves the diversity by employing personalized Determinental Point Process (DPP). DPP has been applied in some recommender systems to improve the diversity and increase the user <a class="link-external link-http" href="http://engagement.However" rel="external noopener nofollow">this http URL</a>, DPP does not take into account the fact that users may have individual propensities to the diversity. To overcome such limitation, our re-ranking model proposes a personalized DPP to model the trade-off between accuracy and diversity for each individual user. We implement and deploy the personalized DPP model on alarge scale industrial recommender system. Experimental results on both offline and online demonstrate the efficiency of our proposed re-ranking model.

How to Diversify any Personalized Recommender? A User-centric Pre-processing approach

Abstract:In this paper, we introduce a novel approach to improve the diversity of Top-N recommendations while maintaining recommendation performance. Our approach employs a user-centric pre-processing strategy aimed at exposing users to a wide array of content categories and topics. We personalize this strategy by selectively adding and removing a percentage of interactions from user profiles. This personalization ensures we remain closely aligned with user preferences while gradually introducing distribution shifts. Our pre-processing technique offers flexibility and can seamlessly integrate into any recommender architecture. To evaluate our approach, we run extensive experiments on two publicly available data sets for news and book recommendations. We test various standard and neural network-based recommender system algorithms. Our results show that our approach generates diverse recommendations, ensuring users are exposed to a wider range of items. Furthermore, leveraging pre-processed data for training leads to recommender systems achieving performance levels comparable to, and in some cases, better than those trained on original, unmodified data. Additionally, our approach promotes provider fairness by facilitating exposure to minority or niche categories.

Abstract:Relevant recommendation is a distinctive recommendation scenario in e-commerce platforms, which provides an extended set of items that are relevant to the trigger item (the item that triggers the relevant recommendation). Different from the general recommendations whose item feeds are diversified, relevant recommendation regards the trigger item as a key component. From one perspective, the trigger item reveals users' current interests and determines the range of the recommendation results. From the other perspective, users may have the mindset to look for items that have directional attribute differences from the trigger item. In this paper, we present an attribute-aware personalized item comparison framework. Under this framework, an item subtraction module is first applied over the trigger item and the candidate item, which calculates their directional difference with consideration of their intrinsic similarity. Then two modules are used to estimate users' preference for this current item pair: one learns the collective preference of all users, and the other learns the current user's personal evolutional preference. Experiments on a CTR prediction task over both a public dataset and an industrial dataset from our shopping app show that the proposed method outperforms the state-of-the-art algorithms and also achieves better generalization ability.

Abstract:In order to increase sales for e-commerce websites and meet customer expectations, recommender systems need to recommend more niche products consumers might like. However, traditional product recommender systems usually aim to improve the recommendation accuracy while overlook the diversity within the recommendation lists. In this paper, firstly we examine the importance of diversity within recommended lists through a psychological survey. Motivated by our observations, we develop a general framework, called DivRec, to improve recommendation diversity without lowering accuracy. Experimental results on an e-commerce dataset demonstrate that our approach outperforms state-of-the-art techniques in terms of both accuracy and diversity.

Abstract:The item details page (IDP) is a web page on an e-commerce website that provides information on a specific product or item listing. Just below the details of the item on this page, the buyer can usually find recommendations for other relevant items. These are typically in the form of a series of modules or carousels, with each module containing a set of recommended items. The selection and ordering of these item recommendation modules are intended to increase discover-ability of relevant items and encourage greater user engagement, while simultaneously showcasing diversity of inventory and satisfying other business objectives. Item recommendation modules on the IDP are often curated and statically configured for all customers, ignoring opportunities for personalization. In this paper, we present a scalable end-to-end production system to optimize the personalized selection and ordering of item recommendation modules on the IDP in real-time by utilizing deep neural networks. Through extensive offline experimentation and online A/B testing, we show that our proposed system achieves significantly higher click-through and conversion rates compared to other existing methods. In our online A/B test, our framework improved click-through rate by 2.48% and purchase-through rate by 7.34% over a static configuration.

Abstract:With the rapid development of e-commerce, the contradiction between the disorder of business information and customer demand is increasingly prominent. This study aims to make e-commerce shopping more convenient, and avoid information overload, by an interactive personalized recommendation system using the hybrid algorithm model. The proposed model first uses various recommendation algorithms to get a list of original recommendation results. Combined with the customer’s feedback in an interactive manner, it then establishes the weights of corresponding recommendation algorithms. Finally, the synthetic formula of evidence theory is used to fuse the original results to obtain the final recommendation products. The recommendation performance of the proposed method is compared with that of traditional methods. The results of the experimental study through a Taobao online dress shop clearly show that the proposed method increases the efficiency of data mining in the consumer coverage, the consumer discovery accuracy and the recommendation recall. The hybrid recommendation algorithm complements the advantages of the existing recommendation algorithms in data mining. The interactive assigned-weight method meets consumer demand better and solves the problem of information overload. Meanwhile, our study offers important implications for e-commerce platform providers regarding the design of product recommendation systems.

Abstract:The need for diversification of recommendation lists manifests in a number of recommender systems use cases. However, an increase in diversity may undermine the utility of the recommendations, as relevant items in the list may be replaced by more diverse ones. In this work we propose a novel method for maximizing the utility of the recommended items subject to the diversity of user's tastes, and show that an optimal solution to this problem can be found greedily. We evaluate the proposed method in two online user studies as well as in an offline analysis incorporating a number of evaluation metrics. The results of evaluations show the superiority of our method over a number of baselines.

Abstract:From e-commerce to music and news, recommender systems are tailored to specific scenarios. While researching generic models applicable to various scenarios is crucial, studying recommendations based on the unique characteristics of a specific and vital scenario holds both research and, more importantly, practical value. In this paper, we focus on store recommendations in the food delivery scenario, which is an intriguing and significant domain with unique behavior patterns and influential factors. First, we offer an in-depth analysis of real-world food delivery data across platforms and countries, revealing that (i) repeat and exploration orders are both noticeable behaviors and (ii) the influences of historical and collaborative situations on repeat and exploration consumption are distinct. Second, based on the observations, we separately design two simple yet effective recommendation models: RepRec for repeat orders and ExpRec for exploration ones. An ensemble module is further proposed to combine recommendations from two models for a unified recommendation list. Finally, experiments are conducted on three datasets spanning three countries across two food delivery platforms. Results demonstrate the superiority of our proposed recommenders on repeat, exploration, and combined recommendation tasks over various baselines. Such simple yet effective approaches will be beneficial for real applications. This work shows that dedicated analyses and methods for domain-specific characteristics are essential for the recommender system studies.
A Reinforcement Learning Approach for Personalized Diversity in Feeds Recommendation.

Abstract:Feeds recommendation has been widely used in various applications, such as e-commerce site, where users can constantly browse products generated by never-ending feeds. It’s important to not only consider instant metrics but also pay more attention to long-term user engagement. In this paper, we focus on optimizing user browsing depth, which represents users’ willingness to stay within the e-commerce feed streams. By analyzing the ranking and re-ranking stages, we find that the re-ranking stage is a suitable phase for maximizing user browsing depth. First, we evaluate the current status of our used re-ranking module and identify that the fixed diversity rule neglects unique propensity to the degree of diversity in each user request. Hence there is a need to personalize diversity in the granularity of user requests. Then, we note that the personalized diversity process of user request granularity can be modelled as a Markov decision process (MDP). Finally, by solving three issues of MDP elements design, acquisition of interaction data, off-policy learning and policy selection, we propose a Personalized Diversity Re-ranking Model in the granularity of user request (PDRM-request) based on reinforcement learning. We conduct offline experiments and deploy the PDRM-request model in a live e-commerce site to perform A/B testing. The results show that the our approach achieves deeper user browsing depth and more diversified recommended lists than the existing baseline.
Optimal Recommendation in the Presense of Comparison Shopping

Abstract:Recommender systems have been widely used by online stores to suggest items of interest to users. These systems often identify a subset of items from a much larger set that best matches the user’s interest. A key concern with existing approaches is over-specialization, which results in returning items that are too similar to each other. Unlike existing solutions that rely on diversity metrics to reduce similarity among recommended items, we propose to use choice probability to measure the overall quality of recommendation lists, which unifies the desire to achieve both relevancy and diversity in generating recommendations. We first define the recommendation problem in the discrete choice setting. We then develop an efficient greedy algorithm that solves the problem to optimum in O(KlogK) time, where K stands for the number of wanted items. Using data from a major travel website, we show that recommendation lists generated by our algorithm outperform existing strong baselines. Sensitivity analysis is also conducted to evaluate the robustness of our solution.

Abstract:Accuracy and diversity have long been considered to be two conflicting goals for recommendations. We point out, however, that as the diversity is typically measured by certain pre-selected item attributes, e.g., category as the most popularly employed one, improved diversity can be achieved without sacrificing recommendation accuracy, as long as the diversification respects the user's preference about the pre-selected attributes. This calls for a fine-grained understanding of a user's preferences over items, where one needs to recognize the user's choice is driven by the quality of the item itself, or the pre-selected attributes of the item. In this work, we focus on diversity defined on item categories. We propose a general diversification framework agnostic to the choice of recommendation algorithms. Our solution disentangles the learnt user representation in the recommendation module into category-independent and category-dependent components to differentiate a user's preference over items from two orthogonal perspectives. Experimental results on three benchmark datasets and online A/B test demonstrate the effectiveness of our solution in improving both recommendation accuracy and diversity. In-depth analysis suggests that the improvement is due to our improved modeling of users' categorical preferences and refined ranking within item categories.

Abstract:Online healthcare communities provide users with various healthcare interventions to promote healthy behavior and improve adherence. When faced with too many intervention choices, however, individuals may find it difficult to decide which option to take, especially when they lack the experience or knowledge to evaluate different options. The choice overload issue may negatively affect users' engagement in health management. In this study, we take a design-science perspective to propose a recommendation framework that helps users to select healthcare interventions. Taking into account that users' health behaviors can be highly dynamic and diverse, we propose a multi-armed bandit (MAB)-driven recommendation framework, which enables us to adaptively learn users' preference variations while promoting recommendation diversity in the meantime. To better adapt an MAB to the healthcare context, we synthesize two innovative model components based on prominent health theories. The first component is a deep-learning-based feature engineering procedure, which is designed to learn crucial recommendation contexts in regard to users' sequential health histories, health-management experiences, preferences, and intrinsic attributes of healthcare interventions. The second component is a diversity constraint, which structurally diversifies recommendations in different dimensions to provide users with well-rounded support. We apply our approach to an online weight management context and evaluate it rigorously through a series of experiments. Our results demonstrate that each of the design components is effective and that our recommendation design outperforms a wide range of state-of-the-art recommendation systems. Our study contributes to the research on the application of business intelligence and has implications for multiple stakeholders, including online healthcare platforms, policymakers, and users.
Beyond Item Dissimilarities: Diversifying by Intent in Recommender Systems

Abstract:Recommender systems that overly focus on short-term engagement prevents users from exploring diverse interests. To tackle this challenge, numerous diversification algorithms have been proposed. These algorithms typically rely on measures of item similarity, aiming to maximize the dissimilarity across items in the final set of recommendations. In this work, we demonstrate the benefits of going beyond item-level similarities by utilizing higher-level user understanding--specifically, user intents that persist across multiple interactions or recommendation sessions--in diversification. Our approach is motivated by the observation that user behaviors on online platforms are largely driven by their underlying intents. Therefore, final recommendations should ensure that a diverse set of intents is accurately represented. While user intent has primarily been studied in the context of search, it is less clear how to incorporate real-time dynamic intent predictions in recommender systems. To address this gap, we develop a probabilistic intent-based whole-page diversification framework for the final stage of a recommender system. Starting with a prior belief of user intents, the proposed framework sequentially selects items for each position based on these beliefs and subsequently updates posterior beliefs about the intents. This approach ensures that different user intents are represented on a page, towards optimizing long-term user experience. We experiment with the intent diversification framework on YouTube. Live experiments on a diverse set of intents show that our framework increases Daily Active Users and overall user enjoyment, validating its effectiveness in facilitating long-term planning. Specifically, it enables users to consistently discover and engage with diverse content that aligns with their underlying intents over time, leading to an improved long-term user experience.

Learning to Personalize Recommendation based on Customers' Shopping Intents

Abstract:Understanding the customers' high level shopping intent, such as their desire to go camping or hold a birthday party, is critically important for an E-commerce platform; it can help boost the quality of shopping experience by enabling provision of more relevant, explainable, and diversified recommendations. However, such high level shopping intent has been overlooked in the industry due to practical challenges. In this work, we introduce Amazon's new system that explicitly identifies and utilizes each customer's high level shopping intents for personalizing recommendations. We develop a novel technique that automatically identifies various high level goals being pursued by the Amazon customers, such as "go camping", and "preparing for a beach party". Our solution is in a scalable fashion (in 14 languages across 21 countries). Then a deep learning model maps each customer's online behavior, e.g. product search and individual item engagements, into a subset of high level shopping intents. Finally, a realtime ranker considers both the identified intents as well as the granular engagements to present personalized intent-aware recommendations. Extensive offline analysis ensures accuracy and relevance of the new recommendations and we further observe an 10% improvement in the business metrics. Abstract:Feed recommendation systems, which recommend a sequence of items for users to browse and interact with, have gained significant popularity in practical applications. In feed products, users tend to browse a large number of items in succession, so the previously viewed items have a significant impact on users' behavior towards the following items. Therefore, traditional methods that mainly focus on improving the accuracy of recommended items are suboptimal for feed recommendations because they may recommend highly similar items. For feed recommendation, it is crucial to consider both the accuracy and diversity of the recommended item sequences in order to satisfy users' evolving interest when consecutively viewing items. To this end, this work proposes a general re-ranking framework named Multi-factor Sequential Re-ranking with Perception-Aware Diversification (MPAD) to jointly optimize accuracy and diversity for feed recommendation in a sequential manner. Specifically, MPAD first extracts users' different scales of interests from their behavior sequences through graph clustering-based aggregations. Then, MPAD proposes two sub-models to respectively evaluate the accuracy and diversity of a given item by capturing users' evolving interest due to the ever-changing context and users' personal perception of diversity from an item sequence perspective. This is consistent with the browsing nature of the feed scenario. Finally, MPAD generates the return list by sequentially selecting optimal items from the candidate set to maximize the joint benefits of accuracy and diversity of the entire list. MPAD has been implemented in Taobao's homepage feed to serve the main traffic and provide services to recommend billions of items to hundreds of millions of users every day.
