Abstract:As one of the most significant components of Intelligent Transportation Systems (ITS), traffic prediction has gained much popularity given its enormous application value in vehicular communications, traffic management, and traffic control. As such, many traffic prediction models have been proposed. The current methods commonly adopt graph convolution networks (GCNs) to capture spatial correlations. GCN-based approaches mainly focus on pair-wise interactions between road vertices (i.e. dyadic relations). However, the interactions between road vertices are not necessarily dyadic, but also can be high-order (i.e., multivariate relations). Further, few existing works focus on how to mine correlations between different types of traffic data. To this end, we develop STGHCN, a spatial-temporal gated hypergraph convolution network, that not only captures pair-wise and high-order spatial patterns between vertices but also characterizes the type-aware traffic data influences. Specifically, we adopt a spatial gated graph convolution and a hypergraph convolution to explore pair-wise and high-order interactions. More importantly, we design a spatial-temporal aware channel attention mechanism to mine hidden patterns between cross-type traffic features. Extensive experiments conducted on four real-world traffic datasets validate the effectiveness of STGHCN, with STGHCN's MAE, RMSE, and MAPE at between 6.91%-10.00%, 5.42%-8.90%, and 2.54%-5.03% lower than the state-of-the-art methods.
GDFormer: A Graph Diffusing Attention Based Approach for Traffic Flow Prediction

Abstract:In this paper, we propose a novel traffic flow prediction approach, called as Graph Diffusing trans-Former (GDFormer). GDFormer is in architecture of transformer, which is composed by the encoder sequence and decoder sequence. both of the encoder sequence and decoder sequence in GDFormer are constituted by the novel designed Graph Diffusing Attention (GDA) module and the auxiliaries. The GDA module utilizes the query-key-value attention to learn the diffusion parameters for each diffusion step, and dynamically updates the adjacency transition, which reflects the dynamically changing traffic flow between the traffic monitors. To verify the efficiency of our approach, we conduct a lot of experiments on two real-world data sets. With a comparison between our approach and the benchmarks, we find that our approach has achieved state of the art performance. Ablation experiments are conducted to illustrate the effectiveness of the key components in the model. Abstract:Traffic information can reflect the operating status of a city, and accurate traffic forecasting is critical in intelligent transportation systems (ITS) and urban planning. However, traffic information has complex nonlinearity and dynamic spatial-temporal dependencies due to human mobility, bringing new traffic forecasting challenges. This paper proposed a graph spatial-temporal transformer network for traffic prediction (GSTTN) to cope with the above problems. Specifically, the proposed framework explores spatial characteristics of the across-road network of traffic information hidden in human behavior patterns via a multi-view graph convolutional network (GCN). Furthermore, the transformer network with a multi-head attention mechanism is adopted to capture the random disturbance in the time series characteristics of traffic information. As a result, these two components can be used to model spatial relations and temporal trends. Finally, we examine real-world datasets, and the experiments show that the proposed framework outperforms the current state-of-the-art baselines.

STGformer: Efficient Spatiotemporal Graph Transformer for Traffic Forecasting

Abstract:Traffic forecasting is a cornerstone of smart city management, enabling efficient resource allocation and transportation planning. Deep learning, with its ability to capture complex nonlinear patterns in spatiotemporal (ST) data, has emerged as a powerful tool for traffic forecasting. While graph neural networks (GCNs) and transformer-based models have shown promise, their computational demands often hinder their application to real-world road networks, particularly those with large-scale spatiotemporal interactions. To address these challenges, we propose a novel spatiotemporal graph transformer (STGformer) architecture. STGformer effectively balances the strengths of GCNs and Transformers, enabling efficient modeling of both global and local traffic patterns while maintaining a manageable computational footprint. Unlike traditional approaches that require multiple attention layers, STG attention block captures high-order spatiotemporal interactions in a single layer, significantly reducing computational cost. In particular, STGformer achieves a 100x speedup and a 99.8\% reduction in GPU memory usage compared to STAEformer during batch inference on a California road graph with 8,600 sensors. We evaluate STGformer on the LargeST benchmark and demonstrate its superiority over state-of-the-art Transformer-based methods such as PDFormer and STAEformer, which underline STGformer's potential to revolutionize traffic forecasting by overcoming the computational and memory limitations of existing approaches, making it a promising foundation for future spatiotemporal modeling tasks.

Abstract:Inter-city highway transportation is significant for urban life. As one of the key functions in intelligent transportation system (ITS), traffic evaluation always plays significant role nowadays, and daily traffic flow prediction still faces challenges at network-wide toll stations. On the one hand, the data imbalance in practice among various locations deteriorates the performance of prediction. On the other hand, complex correlative spatio-temporal factors cannot be comprehensively employed in long-term duration. In this paper, a prediction method is proposed for daily traffic flow in highway domain through spatio-temporal deep learning. In our method, data normalization strategy is used to deal with data imbalance, due to long-tail distribution of traffic flow at network-wide toll stations. And then, based on graph convolutional network, we construct networks in distinct semantics to capture spatio-temporal features. Beside that, meteorology and calendar features are used by our model in the full connection stage to extra external characteristics of traffic flow. By extensive experiments and case studies in one Chinese provincial highway, our method shows clear improvement in predictive accuracy than baselines and practical benefits in business.

Abstract:Accurately predicting traffic flow is paramount for the efficient operation of transportation systems. The key to enhancing prediction accuracy lies in effectively mining the intricate spatio-temporal correlations within traffic flow data. However, traditional traffic flow prediction methods that combine Graph Convolutional Network and Recurrent Neural Network have limitations in capturing comprehensive spatial correlation information and face challenges in modeling long-term temporal dependencies, consequently leading to suboptimal prediction performance. This study proposes a hybrid traffic flow prediction model based on fusion graph convolutional network and enhanced gate recurrent unit. Initially, a fusion graph structure is constructed based on adjacency graph and adaptive graph to better represent the correlations between nodes in the road network. Subsequently, the stacked fusion graph convolution module is utilized to capture multi-level spatial correlations and the enhanced gated recurrent unit is applied to extract multi-scale temporal correlations. In addition, the model integrates the extracted spatio-temporal features with the direct features through residual connection units, and utilizes the fused features for prediction, achieving superior predictive performance. The experimental results from four authentic datasets demonstrate that our proposed model outperforms state-of-the-art baseline models, showcasing an average enhancement of 3% in Mean Absolute Error(MAE), 3.3% in Root Mean Square Error(RMSE), and 2.7% in Mean Absolute Percentage Error(MAPE) across the four datasets.

Abstract:Traffic prediction plays a significant part in creating intelligent cities such as traffic management, urban computing, and public safety. Nevertheless, the complex spatio-temporal linkages and dynamically shifting patterns make it somewhat challenging. Existing mainstream traffic prediction approaches heavily rely on graph convolutional networks and sequence prediction methods to extract complicated spatio-temporal patterns statically. However, they neglect to account for dynamic underlying correlations and thus fail to produce satisfactory prediction results. Therefore, we propose a novel Self-Adaptive Spatio-Temporal Graph Convolutional Network (SASTGCN) for traffic prediction. A self-adaptive calibrator, a spatio-temporal feature extractor, and a predictor comprise the bulk of the framework. To extract the distribution bias of the input in the self-adaptive calibrator, we employ a self-supervisor made of an encoder–decoder structure. The concatenation of the bias and the original characteristics are provided as input to the spatio-temporal feature extractor, which leverages a transformer and graph convolution structures to learn the spatio-temporal pattern, and then applies a predictor to produce the final prediction. Extensive trials on two public traffic prediction datasets (METR-LA and PEMS-BAY) demonstrate that SASTGCN surpasses the most recent techniques in several metrics.

Abstract:Accurate traffic flow prediction is essential to address traffic issues and assist traffic managers make informed decisions in intelligent transportation systems. Extracting potential features from traffic data is challenging due to the complex topology of urban road networks and the time-varying traffic flow. To capture the global spatiotemporal characteristics of traffic flow, we propose a novel model based on graph convolutional networks with a parallel attention network and stacked gated recurrent units (PAGCN-SGRU). First, the parallel attention (PA) network enhances the feature representation of global traffic road nodes and road segments. Then, the graph convolutional networks (GCN) are designed to extract spatial characteristics. Next, the stacked gate recurrent units (SGRU) are employed to capture temporal features. Finally, PAGCN-SGRU discovers global spatiotemporal features for traffic flow prediction. The experimental results demonstrate that the accuracy of PAGCN-SGRU under the SZ-dataset is improved by 9.76 , 72.54 , 5.76 , 16.07 , 2.07 , 1.82 , 3.35 , and 6.59 , respectively, compared to that of HA, ARIMA, SVR, GCN, T-GCN, A3T-GCN, ST-GCN, and DCRNN. In the Los-dataset, the accuracy values increase by 7.11 , 8.94 , 6.66 , 7.77 , 3.43 , 2.45 , 2.28 , and 4.09 , respectively.

Abstract:Traffic flow prediction is an important part of ITS, accurate traffic flow prediction plays a crucial role in the development of ITS. It can not only effectively avoid traffic problems such as traffic congestion, but also provide a database for other complex tasks. With the increase of population and vehicles, the huge amount of traffic data brings a huge challenge to the accuracy of traffic model prediction. Most of the existing methods use some simple spatial-temporal components and static graph structures, and do not distinguish between normal and abnormal traffic flow signals, which is difficult to capture complex temporal and spatial correlations. To solve this problem, we propose a spatial-temporal Transformer with double recurrent graph convolutional cooperative network (STTDGRU) for traffic flow prediction. The model uses the double graph convolutional gated recurrent module based on dynamic graphs to capture the temporal and spatial correlations, and then uses the spatial-temporal Transformer to capture the temporal and spatial correlations in depth, then predicts more accurate traffic flow by integrating multi-level temporal and spatial features. We also use a residual separation superposition mechanism to separate normal and abnormal traffic flow signals and learn the abnormal signals separately. We conduct extensive experiments on four real datasets to demonstrate the effectiveness of the proposed model and its competitiveness with some current methods.

Abstract:Predicting traffic flow is vital for advancing intelligent transportation systems, but achieving precise forecasts remains challenging. To deeply explore the complex and diverse dynamic spatio-temporal correlation of traffic data, this study proposes a multi-information fusion spatio-temporal dynamic graph convolution model for traffic flow prediction. In the model construction, firstly, a dynamic graph generation module is designed to fully capture the complex spatial correlation of the traffic network and model the changing spatio-temporal interaction; secondly, the spatial self-attention mechanism is used to dynamically focus on the spatial relationship between different nodes, and combined with the dynamic graph convolution network to extract the spatial dynamic correlation features of the road network to study deep spatiotemporal information; Finally, existing models rarely consider other traffic information related to traffic flow, and a spatiotemporal information fusion module is designed to enhance the ability of the model to perceive information, thereby improving the performance of traffic flow prediction models. Experiments are conducted on four real traffic datasets using three performance evaluation metrics and 18 baseline models. The results show that the model has higher prediction accuracy.

Abstract:Traffic flow prediction plays a key role in the construction of intelligent transportation system. However, due to its complex spatio-temporal dependence and its uncertainty, the research becomes very challenging. Most of the existing studies are based on graph neural networks that model traffic flow graphs and try to use fixed graph structure to deal with the relationship between nodes. However, due to the time-varying spatial correlation of the traffic network, there is no fixed node relationship, and these methods cannot effectively integrate the temporal and spatial features. This paper proposes a novel temporal-spatial dynamic graph convolutional network (TSADGCN). The dynamic time warping algorithm (DTW) is introduced to calculate the similarity of traffic flow sequence among network nodes in the time dimension, and the spatiotemporal graph of traffic flow is constructed to capture the spatiotemporal characteristics and dependencies of traffic flow. By combining graph attention network and time attention network, a spatiotemporal convolution block is constructed to capture spatiotemporal characteristics of traffic data. Experiments on open data sets PEMSD4 and PEMSD8 show that TSADGCN has higher prediction accuracy than well-known traffic flow prediction algorithms.

Abstract:Abstract Accurate traffic forecasting is more necessary than ever for transportation departments, especially given its significant role in traffic planning, management, and control. However, most existing methods struggle to address complex spatial correlations on road networks, nonlinear temporal dynamics, and difficult long‐term prediction. This article proposes a novel spatial temporal graph gated transformer (STGGT) to overcome these challenges. The suggested model differs from Google's transformer because it uses a hybrid architecture that integrates graph convolutional networks (GCNs), attention, and gated recurrent units (GRUs) instead of solely relying on attention. Specifically, STGGT uses GCNs to extract spatial dependencies, utilizes attention and GRUs to extract temporal dependencies, and handle long‐term prediction. Experiments indicate that STGGT outperforms the state‐of‐the‐art baseline models on two real‐world traffic datasets of 9%–40%. The proposed model offers a promising solution for accurate traffic forecasting, simultaneously addressing the challenges of complex spatial correlations, nonlinear temporal dynamics, and long‐term prediction.

Dynamic Graph Convolutional Network with Attention Fusion for Traffic Flow Prediction

Abstract:Accurate and real-time traffic state prediction is of great practical importance for urban traffic control and web mapping services. With the support of massive data, deep learning methods have shown their powerful capability in capturing the complex spatialtemporal patterns of traffic networks. However, existing approaches use pre-defined graphs and a simple set of spatial-temporal components, making it difficult to model multi-scale spatial-temporal dependencies. In this paper, we propose a novel dynamic graph convolution network with attention fusion to tackle this gap. The method first enhances the interaction of temporal feature dimensions, and then it combines a dynamic graph learner with GRU to jointly model synchronous spatial-temporal correlations. We also incorporate spatial-temporal attention modules to effectively capture longrange, multifaceted domain spatial-temporal patterns. We conduct extensive experiments in four real-world traffic datasets to demonstrate that our method surpasses state-of-the-art performance compared to 18 baseline methods.

Abstract:Extensive traffic flow data are received from the loop detector networks every second, which requires us to develop an effective and efficient algorithm to predict future traffic flow. However, dynamic traffic conditions on a road are not just influenced by sequential patterns in the temporal dimension, but also by other roadways in the spatial dimension. Although many successful models have been developed in previous studies to forecast future traffic flows, most of them have shortcomings in modeling spatial and temporal dependencies. In this article, we focus on spatial-temporal factors and propose a new adaptive spatial-temporal transformer graph network (ASTTGN) to improve the accuracy of traffic forecasting by jointly modeling the spatial-temporal information of road networks. Specifically, we propose an adaptive spatial-temporal transformer module, which contains two developed adaptive transformer modules for capturing dynamic spatial dependence and temporal dependence across multiple time steps, respectively. Finally, feature fusion is performed through a gated feature aggregation layer to simulate the effect of complex spatial-temporal factors on traffic conditions. In particular, the multihead attention mechanism employed by the transformer can effectively explore the potential spatial-temporal dependence patterns in different subspaces. Experimental results on two real-world traffic data sets demonstrate the superiority of the proposed model compared to existing techniques.

Abstract:Accurate prediction of traffic flow plays an important role in maintaining traffic order and traffic safety, which is a key task in the application of intelligent transportation systems (ITS). However, the urban road network has complex dynamic spatial correlation and nonlinear temporal correlation, and achieving accurate traffic flow prediction is a highly challenging task. Traditional methods use sensors deployed on roads to construct the spatial structure of the road network and capture spatial information by graph convolution. However, they ignore that the spatial correlation between nodes is dynamically changing, and using a fixed adjacency matrix cannot reflect the real road spatial structure. To overcome these limitations, this paper proposes a new spatial-temporal deep learning model: gated fusion adaptive graph neural network (GFAGNN). GFAGNN first extracts long-term dependencies on raw data through stacking expansion causal convolution, Then the spatial features of the dynamics are learned by adaptive graph attention network and adaptive graph convolutional network respectively, Finally the fused information is passed through a lightweight channel attention to extract temporal features. The experimental results on two public data sets show that our model can effectively capture the spatiotemporal correlation in traffic flow prediction. Compared with GWNET-conv model on METR-LA dataset, the three indexes in the 60-minute task prediction improved by 2.27%,2.06% and 2.13%, respectively.

Abstract:Traffic forecasting is significant for establishing intelligent traffic systems. However, the complex spatial-temporal relationships of traffic flow data make it challenging. Despite some studies investigating this problem, capturing complex spatial structures and learning the temporal dependence of the long-term prediction are still challenges that need to be addressed. In this paper, we propose a novel attention-based spatial-temporal graph transformer (ASTGT) model to solve the traffic flow forecasting problem. ASTGT primarily consists of two independent components: temporal encoder and spatial-temporal decoder. Precisely, in temporal encoder, we capture the temporal dynamics of traffic data through the self-attention mechanism. The traffic flow data with long-term periodic dependence are also integrated. Moreover, spatial-temporal decoder superimposes the gated spatial graph convolution block to acquire both temporal and spatial relationships at the same time. Extensive experiments are conducted on PEMS04 and PEMS08 datasets from the Caltrans Performance Measurement System. The results show that our proposed ASTGT model outperforms the state-of-the-art baselines.

Navigating Spatio-Temporal Heterogeneity: A Graph Transformer Approach for Traffic Forecasting

Abstract:Traffic forecasting has emerged as a crucial research area in the development of smart cities. Although various neural networks with intricate architectures have been developed to address this problem, they still face two key challenges: i) Recent advancements in network designs for modeling spatio-temporal correlations are starting to see diminishing returns in performance enhancements. ii) Additionally, most models do not account for the spatio-temporal heterogeneity inherent in traffic data, i.e., traffic distribution varies significantly across different regions and traffic flow patterns fluctuate across various time slots. To tackle these challenges, we introduce the Spatio-Temporal Graph Transformer (STGormer), which effectively integrates attribute and structure information inherent in traffic data for learning spatio-temporal correlations, and a mixture-of-experts module for capturing heterogeneity along spaital and temporal axes. Specifically, we design two straightforward yet effective spatial encoding methods based on the graph structure and integrate time position encoding into the vanilla transformer to capture spatio-temporal traffic patterns. Additionally, a mixture-of-experts enhanced feedforward neural network (FNN) module adaptively assigns suitable expert layers to distinct patterns via a spatio-temporal gating network, further improving overall prediction accuracy. Experiments on real-world traffic datasets demonstrate that STGormer achieves state-of-the-art performance.

Abstract:Traffic prediction is a core problem in the intelligent transportation system and has broad applications in the transportation management and planning, and the main challenge of this field is how to efficiently explore the spatial and temporal information of traffic data. Recently, various deep learning methods, such as convolution neural network (CNN), have shown promising performance in traffic prediction. However, it samples traffic data in regular grids as the input of CNN, thus it destroys the spatial structure of the road network. In this paper, we introduce a graph network and propose an optimized graph convolution recurrent neural network for traffic prediction, in which the spatial information of the road network is represented as a graph. Additionally, distinguishing with most current methods using a simple and empirical spatial graph, the proposed method learns an optimized graph through a data-driven way in the training phase, which reveals the latent relationship among the road segments from the traffic data. Lastly, the proposed method is evaluated on three real-world case studies, and the experimental results show that the proposed method outperforms state-of-the-art traffic prediction methods.

Abstract:With the rapid development of economy, the sharp increase in the number of urban cars and the backwardness of urban road construction lead to serious traffic congestion of urban roads. Many scholars have tried their best to solve this problem by predicting traffic congestion. Some traditional models such as linear models and nonlinear models have been proved to have a good prediction effect. However, with the increasing complexity of urban traffic network, these models can no longer meet the higher demand of congestion prediction without considering more complex comprehensive factors, such as the spatio-temporal correlation information between roads. In this paper, we propose a traffic congestion index and devise a new traffic congestion prediction model spatio-temporal transformer (STTF) based on transformer, a deep learning model. The model comprehensively considers the traffic speed of road segments, road network structure, the spatio-temporal correlation between road sections and so on. We embed temporal and spatial information into the model through the embedding layer for learning, and use the spatio-temporal attention module to mine the hidden spatio-temporal information within the data to improve the accuracy of traffic congestion prediction. Experimental results based on real-world datasets demonstrate that the proposed model significantly outperforms state-of-the-art approaches.

Abstract:Traffic flow prediction, which provides dynamic data support for intelligent transportation systems, has always been a topic of great interest. Accurate prediction of traffic flow is vital for optimizing traffic management and planning and improving traffic efficiency. Existing traffic flow prediction models usually consider only a single influencing factor when modeling spatial-temporal correlation and fail to comprehensively consider the multiscale factors corresponding to each module, resulting in incomplete spatial-temporal modeling and thus affecting prediction accuracy. For this reason, this paper proposes a spatial-temporal multifactor fusion graph neural network (STMFGNN), which aims to characterize spatial-temporal features more comprehensively. First, in the spatial feature extraction module, we parallelly utilize dynamic similarity graphs and static adjacency graphs to perform graph convolution and introduce the gated fusion module to self-learn the dynamic influence weight so that our model can integrate the information of global hidden knowledge and local prior knowledge and capture the multiscale spatial dependencies between nodes. Second, the model combines gated tanh unit convolution with a multireceptive field and gated recurrent units in the temporal feature extraction module. Similarly, it utilizes the gated fusion module to adaptively and dynamically adjust the importance weights of the two components. This enables the acquisition of multiscale temporal dependency information at both short-term and long-term levels. In addition, we employ an improved generative adversarial imputation network for incomplete traffic flow data. The experimental results on four real-world datasets show that our proposed method consistently outperforms other baseline models, achieving state-of-the-art performance.
