Abstract:Recently, deep learning approach has achieved promising results in various fields of computer vision. In this paper, a new framework called Hierarchical Depth Motion Maps (HDMM) + 3 Channel Deep Convolutional Neural Networks (3ConvNets) is proposed for human action recognition using depth map sequences. Firstly, we rotate the original depth data in 3D pointclouds to mimic the rotation of cameras, so that our algorithms can handle view variant cases. Secondly, in order to effectively extract the body shape and motion information, we generate weighted depth motion maps (DMM) at several temporal scales, referred to as Hierarchical Depth Motion Maps (HDMM). Then, three channels of ConvNets are trained on the HDMMs from three projected orthogonal planes separately. The proposed algorithms are evaluated on MSRAction3D, MSRAction3DExt, UTKinect-Action and MSRDailyActivity3D datasets respectively. We also combine the last three datasets into a larger one (called Combined Dataset) and test the proposed method on it. The results show that our approach can achieve state-of-the-art results on the individual datasets and without dramatical performance degradation on the Combined Dataset.

Action Recognition By Learning Deep Multi-Granular Spatio-Temporal Video Representation

Abstract:Recognizing actions in videos is a challenging task as video is an information-intensive media with complex variations. Most existing methods have treated video as a flat data sequence while ignoring the intrinsic hierarchical structure of the video content. In particular, an action may span different granularities in this hierarchy including, from small to large, a single frame, consecutive frames (motion), a short clip, and the entire video. In this paper, we present a novel framework to boost action recognition by learning a deep spatio-temporal video representation at hierarchical multi granularity. Specifically, we model each granularity as a single stream by 2D (for frame and motion streams) or 3D (for clip and video streams) convolutional neural networks (CNNs). The framework therefore consists of multi-stream 2D or 3D CNNs to learn both the spatial and temporal representations. Furthermore, we employ the Long Short-Term Memory (LSTM) networks on the frame, motion, and clip streams to exploit long-term temporal dynamics. With a softmax layer on the top of each stream, the classification scores can be predicted from all the streams, followed by a novel fusion scheme based on the multi-granular score distribution. Our networks are learned in an end-to-end fashion. On two video action benchmarks of UCF101 and HMDB51, our framework achieves promising performance compared with the state-of-the-art.
Depth2Action: Exploring Embedded Depth for Large-Scale Action Recognition

Abstract:This paper performs the first investigation into depth for large-scale human action recognition in video where the depth cues are estimated from the videos themselves. We develop a new framework called depth2action and experiment thoroughly into how best to incorporate the depth information. We introduce spatio-temporal depth normalization (STDN) to enforce temporal consistency in our estimated depth sequences. We also propose modified depth motion maps (MDMM) to capture the subtle temporal changes in depth. These two components significantly improve the action recognition performance. We evaluate our depth2action framework on three large-scale action recognition video benchmarks. Our model achieves state-of-the-art performance when combined with appearance and motion information thus demonstrating that depth2action is indeed complementary to existing approaches.

Abstract:Detecting actions in videos, particularly within cluttered scenes, poses significant challenges due to the limitations of 2D frame analysis from a camera perspective. Unlike human vision, which benefits from 3D understanding, recognizing actions in such environments can be difficult. This research introduces a novel approach integrating 3D features and depth maps alongside RGB features to enhance action recognition accuracy. Our method involves processing estimated depth maps through a separate branch from the RGB feature encoder and fusing the features to understand the scene and actions comprehensively. Using the Side4Video framework and VideoMamba, which employ CLIP and VisionMamba for spatial feature extraction, our approach outperformed our implementation of the Side4Video network on the Something-Something V2 dataset. Online Robust Action Recognition Based on a Hierarchical Model

Abstract:With the strong demand for human machine interaction, action recognition has attracted more and more attention in recent years. Traditional video-based approaches are very sensitive to background activity, and also lack the ability to discriminate complex 3D motion. With the emergence and development of commercial depth cameras, action recognition based on 3D skeleton joints is becoming more and more popular. However, a skeleton-based approach is still very challenging because of the large variation in human actions and temporal dynamics. In this paper, we propose a hierarchical model for action recognition. To handle confusing motions in a large feature space, a motion-based grouping method is first proposed, which can efficiently assign each video a group label, and then for each group, a pre-trained classifier is used for frame-labeling. Unlike previous methods, we adopt a bottom-up approach that first performs action recognition for each frame. The final action label is obtained by fusing the classification to its frames, with the effect of each frame being adaptively adjusted based on its local properties. The proposed method is evaluated using two challenge datasets captured by a Kinect. Experiments show that our method can perform more robustly than state-of-the-art approaches.

Abstract:Dynamic imaging is a recently proposed action description paradigm for simultaneously capturing motion and temporal evolution information, particularly in the context of deep convolutional neural networks (CNNs). Compared with optical flow for motion characterization, dynamic imaging exhibits superior efficiency and compactness. Inspired by the success of dynamic imaging in RGB video, this study extends it to the depth domain. To better exploit three-dimensional (3D) characteristics, multi-view dynamic images are proposed. In particular, the raw depth video is densely projected with respect to different virtual imaging viewpoints by rotating the virtual camera within the 3D space. Subsequently, dynamic images are extracted from the obtained multi-view depth videos and multi-view dynamic images are thus constructed from these images. Accordingly, more view-tolerant visual cues can be involved. A novel CNN model is then proposed to perform feature learning on multi-view dynamic images. Particularly, the dynamic images from different views share the same convolutional layers but correspond to different fully connected layers. This is aimed at enhancing the tuning effectiveness on shallow convolutional layers by alleviating the gradient vanishing problem. Moreover, as the spatial occurrence variation of the actions may impair the CNN, an action proposal approach is also put forth. In experiments, the proposed approach can achieve state-of-the-art performance on three challenging datasets.

Abstract:This paper presents a new framework for human action recognition from depth sequences. An effective depth feature representation is developed based on the fusion of 2D and 3D auto-correlation of gradients features. Specifically, depth motion maps (DMMs) are first employed to transform a depth sequence into three images capturing shape and motion cues. A feature extraction method utilizing spatial and orientational auto-correlations of image local gradients is introduced to extract features from DMMs. Space-time auto-correlation of gradients features are also extracted from depth sequences as complementary features to cope with the temporal information loss in the DMMs generation. Each set of features is used as input to two extreme learning machine classifiers to generate probability outputs. A weighted fusion strategy is proposed to assign different weights to the classifier probability outputs associated with different features, thereby providing more flexibility in the final decision making. The proposed method is evaluated on two depth action datasets (MSR Action 3D and MSR Gesture 3D) and obtains the state-of-the-art recognition performance (94.87 % for the MSR Action 3D and 98.50 % for the MSR Gesture 3D).

Abstract:In the field of human action recognition (HAR), two-stream models have been widely employed. In recent years, traditional two-stream network models have disregarded the interframe sequence characteristics of video, resulting in a decrease in model robustness when local sequence information and long-term motion information interact. In light of this, a novel three-stream neural network is proposed by combining the long-term and short-term characteristics of a frame sequence with spatio-temporal information. Initially, the optical flow sequence image frames and RGB image frames in the video are extracted, the optical flow motion information and image space information in the video is obtained, the corresponding time network and space network are entered, and the spatial information is entered into the sequence feature processing network; the three networks are then pretrained. At the conclusion of training, the operation of feature extraction is executed, the features are incorporated with the parallel fusion algorithm by adding weights, and the behavior categories are classified using Multi-Layer Perception. Experimental results on the UCF11, UCF50, and HMDB51 datasets demonstrate that our model effectively integrates the spatial-temporal and frame-sequence information of human actions, resulting in a significant improvement in recognition accuracy. Its classification accuracy on the three datasets was 99.17%, 97.40%, and 96.88%, respectively, significantly enhancing the generalization capability and validity of conventional two-stream or three-stream models.

Abstract:The goal of human action recognition is to identify and understand the actions of people in videos and export corresponding tags. In addition to spatial correlation existing in 2D images, actions in a video also own the attributes in temporal domain. Due to the complexity of human actions, e.g., the changes of perspectives, background noises, and others will affect the recognition. In order to solve these thorny problems, three algorithms are designed and implemented in this paper. Based on convolutional neural networks (CNN), Two-Stream CNN, CNN+LSTM, and 3D CNN are harnessed to identify human actions in videos. Each algorithm is explicated and analyzed on details. HMDB-51 dataset is applied to test these algorithms and gain the best results. Experimental results showcase that the three methods have effectively identified human actions given a video, the best algorithm thus is selected.

Abstract:This work presents a real-time human action recognition system that uses depth map sequence as input. The system contains the segmentation of human, the action modeling based on 3D shape context and the action graph algorithm. We effectively solve the problem of segmenting human from complex and cluttered scenes by combing a novel quadtree split-and-merge method and the codebook background modeling algorithm. We aims at recognizing actions that are used in games and interactions, especially complex actions that contain foot motion and body heave. By expanding the shape context descriptor into 3D space, we obtain translation and scale invariant features and get rid of normalization error, which is a common problem of real-life applications. Experiments in various scenarios demonstrate the high speed and excellent performance of our procedure.
A very deep sequences learning approach for human action recognition

Abstract:Human action recognition is a popular study in computer vision. The most difficult challenge is capturing the movement features of image sequences or videos. In recent years, deep convolutional networks have achieved great success in many image classification and recognition tasks. But in videos interpretation tasks, the deep-learning has not done well. There were [18, 19] earlier models which were built on convolutional networks for human action recognition tasks. We propose an approach based on CNNs and RNN-like models which have abilities to extract spatial and temporal features both, a CNN model can get static scores, a LSTM or GRU layer which gets dynamic class scores of human action. In another side, compared to a two-stream ConvNet [18, 24], we do not need an optical-flow CNN stream that saves us considerable time, RNN-like models just need a few hours to get convergence. And, we have achieved a quite remarkable performance. © Springer International Publishing Switzerland 2016.

Abstract:Single modality action recognition on RGB or depth sequences has been extensively explored recently. It is generally accepted that each of these two modalities has different strengths and limitations for the task of action recognition. Therefore, analysis of the RGB+D videos can help us to better study the complementary properties of these two types of modalities and achieve higher levels of performance. In this paper, we propose a new deep autoencoder based shared-specific feature factorization network to separate input multimodal signals into a hierarchy of components. Further, based on the structure of the features, a structured sparsity learning machine is proposed which utilizes mixed norms to apply regularization within components and group selection between them for better classification performance. Our experimental results show the effectiveness of our cross-modality feature analysis framework by achieving state-of-the-art accuracy for action classification on five challenging benchmark datasets.

Skeleton-Indexed Deep Multi-Modal Feature Learning for High Performance Human Action Recognition

Abstract:This paper presents a new framework for action recognition with multi-modal data. A skeleton-indexed feature learning procedure is developed to further exploit the detailed local features from RGB and optical flow videos. In particular, the proposed framework is built based on a deep Convolutional Network (ConvNet) and a Recurrent Neural Network (RNN) with Long Short Term Memory (LSTM). A skeleton-indexed transform layer is designed to automatically extract visual features around key joints, and a part-aggregated pooling is developed to uniformly regulate the visual features from different body parts and actors. Besides, several fusion schemes are explored to take advantage of multi-modal data. The proposed deep architecture is end-to-end trainable and can better incorporate different modalities to learn effective feature representations. Quantitative experiment results on two datasets, the NTU RGB+D dataset and the MSR dataset, demonstrate the excellent performance of our scheme over other state-of-the-arts. To our knowledge, the performance obtained by the proposed framework is currently the best on the challenging NTU RGB+D dataset.

Abstract:Video analysis is an important branch of computer vision due to its wide applications, ranging from video surveillance, video indexing, and retrieval to human computer interaction. All of the applications are based on a good video representation, which encodes video content into a feature vector with fixed length. Most existing methods treat video as a flat image sequence, but from our observations we argue that video is an information-intensive media with intrinsic hierarchical structure, which is largely ignored by previous approaches. Therefore, in this work, we represent the hierarchical structure of video with multiple granularities including, from short to long, single frame, consecutive frames (motion), short clip, and the entire video. Furthermore, we propose a novel deep learning framework to model each granularity individually. Specifically, we model the frame and motion granularities with 2D convolutional neural networks and model the clip and video granularities with 3D convolutional neural networks. Long Short-Term Memory networks are applied on the frame, motion, and clip to further exploit the long-term temporal clues. Consequently, the whole framework utilizes multi-stream CNNs to learn a hierarchical representation that captures spatial and temporal information of video. To validate its effectiveness in video analysis, we apply this video representation to action recognition task. We adopt a distribution-based fusion strategy to combine the decision scores from all the granularities, which are obtained by using a softmax layer on the top of each stream. We conduct extensive experiments on three action benchmarks (UCF101, HMDB51, and CCV) and achieve competitive performance against several state-of-the-art methods.
3D Action Recognition Using Multi-Temporal Depth Motion Maps and Fisher Vector

Abstract:This paper presents an effective local spatio-temporal descriptor for action recognition from depth video sequences. The unique property of our descriptor is that it takes the shape discrimination and action speed variations into account, intending to solve the problems of distinguishing different pose shapes and identifying the actions with different speeds in one goal. The entire algorithm is carried out in three stages. In the first stage, a depth sequence is divided into temporally overlapping depth segments which are used to generate three depth motion maps (DMMs), capturing the shape and motion cues. To cope with speed variations in actions, multiple frame lengths of depth segments are utilized, leading to a multitemporal DMMs representation. In the second stage, all the DMMs are first partitioned into dense patches. Then, the local binary patterns (LBP) descriptor is exploited to characterize local rotation invariant texture information in those patches. In the third stage, the Fisher kernel is employed to encode the patch descriptors for a compact feature representation, which is fed into a kernel-based extreme learning machine classifier. Extensive experiments on the public MSRAction3D, MSRGesture3D and DHA datasets show that our proposed method outperforms state-of-the-art approaches for depth-based action recognition.

Abstract:Recently, deep convolutional networks (ConvNets) have achieved remarkable progress for action recognition in videos. Most existing deep frameworks treat a video as an unordered frame sequence, and make a prediction by averaging the output of single RGB image, or stacked optical flow field. However, within a video, complex actions may consist of several atomic actions carried out in a sequential manner during its temporal range. To address this issue, we propose a deep learning framework, sequential segment networks (SSN), to model video-level temporal structures in videos. We get several short video snippets by a sparse temporal sampling strategy, and then concatenate the output of ConvNets learned from short snippets; finally, the concatenated consensus vector is fed into a fully connected layer to learn its temporal structure. The sparse sampling strategy and video-level structure enable an efficient and effective training process for SSNs. Extensive empirical studies demonstrate that action recognition performance can be significantly improved by mining temporal structures, and our approach achieves state-of-the-art performance on UCF101 and HMDB51 datasets.
Complex Human Action Recognition Using a Hierarchical Feature Reduction and Deep Learning-Based Method

Abstract:Abstract Automated human action recognition is one of the most attractive and practical research fields in computer vision. In such systems, the human action labelling is based on the appearance and patterns of the motions in the video sequences; however, majority of the existing research and most of the conventional methodologies and classic neural networks either neglect or are not able to use temporal information for action recognition prediction in a video sequence. On the other hand, the computational cost of a proper and accurate human action recognition is high. In this paper, we address the challenges of the preprocessing phase, by an automated selection of representative frames from the input sequences. We extract the key features of the representative frame rather than the entire features. We propose a hierarchical technique using background subtraction and HOG, followed by application of a deep neural network and skeletal modelling method. The combination of a CNN and the LSTM recursive network is considered for feature selection and maintaining the previous information; and finally, a Softmax-KNN classifier is used for labelling the human activities. We name our model as “Hierarchical Feature Reduction & Deep Learning” -based action recognition method, or HFR-DL in short. To evaluate the proposed method, we use the UCF101 dataset for the benchmarking which is widely used among researchers in the action recognition research field. The dataset includes 101 complicated activities in the wild. Experimental results show a significant improvement in terms of accuracy and speed in comparison with eight state-of-the-art methods.
Fast and Reliable Human Action Recognition in Video Sequences by Sequential Analysis

Abstract:Human action recognition from video sequences is a challenging topic in computer vision research. In recent years, many studies have explored the use of deep learning representations to consistently improve the analysis accuracy. Meanwhile, designing a fast and reliable framework is becoming increasingly important given the exponential growth of video data collected for many purposes (e.g. public security, entertainment, and early medical diagnosis etc.). In order to design a more efficient automatic human action annotation method, the sequential probability ratio test, one of the classical statistical sampling scheme, is adapted to solve a multi-classes hypothesis test problem in our work. With the proposed algorithm, the computational cost is reduced significantly without sacrificing the performance of the underlying system. The experimental results based on the UCF101 data set demonstrated the efficiency of the framework compared to the fixed sampling scheme.

Abstract:Depth motion maps (DMMs) have shown effectiveness in human action recognition, however, they lose the temporal information and suffer from intra-class variations caused by action speed variations. To address these challenges, we propose a novel method for human action recognition. Firstly, Adaptive Hierarchical Depth Motion Maps (AH-DMMs) are calculated over temporal hierarchical windows of video sequences to capture the temporal information. Moreover, adaptive windows and steps are employed to ensure that AH-DMMs are robust to motion speed variations. Then, Gabor filter is adopted to encode the texture information of AH-DMMs, generating compact and discriminative action representations. Finally, the representations serve as the input of collaborative representation classifier (CRC). Experimental results on public benchmark MSRAction3D dataset and DHA dataset demonstrate the superiority of the proposed method over the state-of-the-art depth-based action recognition approaches.
DB-LSTM: Densely-connected Bi-directional LSTM for Human Action Recognition

Abstract:Although deep learning has achieved promising progress recently, action recognition remains a challenging task, due to cluttered backgrounds, diverse scenes, occlusions, viewpoint variations and camera motions. In this paper, we propose a novel deep learning model to capture the spatial and temporal patterns of human actions from videos. Sample representation learner is proposed to extract the video-level temporal feature, which combines the sparse temporal sampling and long-range temporal learning to form an efficient and effective training strategy. To boost the effectiveness and robustness of modeling long-range action recognition, a Densely-connected Bi-directional LSTM (DB-LSTM) network is novelly proposed to model the visual and temporal associations in both forward and backward directions. They are stacked and integrated with the dense skip-connections to improve the capability of temporal pattern modeling. Two modalities from appearance and motion are integrated with a fusion module to further improve the performance. Experiments conducted on two benchmark datasets, UCF101 and HMDB51, demonstrate that the proposed DB-LSTM model achieves promising performance, which outperforms the state-of-the-art approaches for action recognition.
