Abstract:The model parameters of the lithium-ion battery are of great importance to model-based battery state estimation methods. The fact that parameters change in different rates with operation temperature, state of charge (SOC), state of health (SOH) and other factors calls for an online parameter identification algorithm that can track different dynamic characters of the parameters. In this paper, a novel multiple forgetting factor recursive least square (MFFRLS) algorithm was proposed. Forgetting factors were assigned to each parameter, allowing the algorithm to capture the different dynamics of the parameters. Particle swarm optimization (PSO) was utilized to determine the optimal forgetting factors. A state of the art SOC estimator, known as the unscented Kalman filter (UKF), was combined with the online parameter identification to create an accurate estimation of SOC. The effectiveness of the proposed method was verified through a driving cycle under constant temperature and three different driving cycles under varied temperature. The single forgetting factor recursive least square (SFFRLS)-UKF and UKF with fixed parameter were also tested for comparison. The proposed MFFRLS-UKF method obtained an accurate estimation of SOC especially when the battery was running in an environment of changing temperature.

Abstract:The state of charge (SOC) and the state of health (SOH) are the two most important indexes of batteries. However, they are not measurable with transducers and must be estimated with mathematical algorithms. A precise model and accurate available battery capacity are crucial to the estimation results. An improved speed adaptive velocity particle swarm optimization algorithm (SAVPSO) based on the Thevenin model is used for online parameter identification, which is used with an unscented Kalman filter (UKF) to estimate the SOC. In order to achieve the cyclic update of the SOH, the concept of degree of polarization (DOP) is proposed. The cyclic update of available capacity is thus obtainable to conversely promote the estimation accuracy of the SOC. The estimation experiments in the whole aging process of batteries show that the proposed method can enhance the SOC estimation accuracy in the full battery life cycle with the cyclic update of the SOH, even in cases of operating aged batteries and under complex operating conditions.

Abstract:With the continuous development of electric vehicles and renewable energy, the rapid and accurate estimation of the State of Charge (SOC) of lithium batteries is crucial for energy storage applications. Traditional Open Circuit Voltage (OCV) measurements, which require prolonged battery rest, are not applicable during battery operation. Therefore, Ampere-Hour Integration is commonly adopted to estimate the battery SOC in real-time during charging and discharging processes. However, this method is prone to cumulative errors, making it challenging to accurately estimate SOC during prolonged battery operation. To address this issue, an adaptive SOC estimation method based on online OCV calibration is proposed in this paper. By establishing the equivalent circuit model (ECM) and combining the experimental test data, the functional relationship between the calibration voltage and the battery resting time is obtained to compensate for the terminal voltage measurement error caused by the battery polarization reaction. Then by using the calibrated OCV, combined with the OCV-SOC relationship obtained from the experimental test, the difference fitting method is used to realize the OCV-SOC online calibration. Based on the SOC estimation results after online OCV calibration, the K-value adaptive mathematical model is established to correct the accumulated error during Ampere-hour integration. Experimental validation and simulation analysis demonstrate the effectiveness of the proposed method in compensating for OCV measurement errors caused by battery polarization and reducing cumulative errors in Ampere-hour integration.

Abstract:Underwater vehicles are important mobile platforms used for ocean exploration. However, temperature changes along the ocean depth are rapid and complex, making it difficult to estimate the SOC (state of charge). Besides, the EKF method, which is used widely for SOC estimation, ignores the higher-order terms of Taylor expansion, which may produce large truncation errors. To address this problem, this paper proposed a SOC estimation method based on the extended Kalman filter and regularised extreme learning machine (EKF-RELM). First, the relationship between model parameters and temperature is explored. Then the EKF is applied to estimate the value of SOC and the RELM is used ultimately to revise the estimated value. Offline experiments were conducted to assess the performance of the EKF-RELM method compared with the EKF method under different conditions. The estimation error of EKF-RELM was less than that of EKF under variable temperature and load conditions. Finally, trials were performed in Qiandao Lake, and the maximum error (ME) in the SOC estimation was found to be less than 1.67%.

Abstract:With the increase in the amount of actual operating data on electric vehicles, how to analyze and process useful information from existing battery charging and discharging data and apply it to subsequent state estimation is worthy of in-depth thinking and practice by researchers. This article proposes a collaborative estimation architecture for SOC and SOH based on the 1RC equivalent circuit model, recursive least squares, and adaptive extended Kalman filtering algorithms (AEKF), which combine offline data processing with online applications. By applying offline data processing, OCV–SOC polynomial fitting and average polarization resistance were determined, which reduced the time required for basic data measurement and improved the accuracy of model parameter identification, while a recursive estimation combining micro- and macro-time-scales of AEKF was used for the online real-time estimation of the SOC and actual available capacity of batteries, in order to eliminate interference from measurement and process noise. The results of the simulated and experimental data validation indicate that the proposed algorithm is applicable to the lithium-ion batteries studied in this paper, the average SOC deviation is less than 1.5%, the maximum deviation is less than 2.02%, and the SOH estimation deviation is less than 1% under different driving conditions in the multi-temperature range. This study lays the foundation for further utilizing offline data and improving SOC and SOH collaborative estimation algorithms.

Abstract:An accurate state of charge (SOC) estimation in battery management systems (BMS) is of crucial importance to guarantee the safe and effective operation of automotive batteries. However, the BMS consistently suffers from inaccuracy of SOC estimation. Herein, we propose a SOC estimation approach with both high accuracy and robustness based on an improved extended Kalman filter (IEKF). An equivalent circuit model is established, and the simulated annealing-particle swarm optimization (SA-PSO) algorithm is used for offline parameter identification. Furthermore, improvements have been made with noise adaptation, a fading filter and a linear-nonlinear filtering based on the traditional EKF method, and rigorous mathematical proof has been carried out accordingly. To deal with model mismatch, online parameter identification is achieved by a dual Kalman filter. Finally, various experiments are performed to validate the proposed IEKF. Experimental results show that the IEKF algorithm can reduce the error to 2.94% under dynamic stress test conditions, and robustness analysis is verified with noise interference, hence demonstrating its practicability for extending to state estimation of battery packs applied in real-world operating conditions.

Abstract:Real-time estimation of the state of charge (SOC) of the battery is a crucial need in the growing fields of plug-in hybrid electric vehicles and smart grid applications. The accuracy of the estimation algorithm directly depends on the accuracy of the model used to describe the characteristics of the battery. Considering a resistance-capacitance (RC)-equivalent circuit to model the battery dynamics, we use a piecewise linear approximation with varying coefficients to describe the inherently nonlinear relationship between the open-circuit voltage (V-OC) and the SOC of the battery. Several experimental test results on lithium (Li)-polymer batteries show that not only do the V-OC-SOC relationship coefficients vary with the SOC and charging/discharging rates but also the RC parameters vary with them as well. The moving window least squares parameter-identification technique was validated by both data obtained from a simulated battery model and experimental data. The necessity of updating the parameters is evaluated using observers with updating and nonupdating parameters. Finally, the SOC coestimation method is compared with the existing well-known SOC estimation approaches in terms of performance and accuracy of estimation.

Abstract:Accurate state of charge (SOC) estimation of traction batteries plays a crucial role in energy and safety management for electric vehicles. Existing studies focus primarily on cell battery SOC estimation. However, numerical instability and divergence problems might occur for a large-size lithium-ion battery pack consisting of many cells. This paper proposes a high-performance online model identification and SOC estimation method based on an adaptive square root unscented Kalman filter (ASRUKF) and an improved forgetting factor recursive least squares (IFFRLS) for vehicle-level traction battery packs. The model parameters are identified online through the IFFRLS, where the conventional method might encounter numerical stability problems. By updating the square root of the covariance matrix, the divergence problem in the traditional unscented Kalman filter is solved in the ASRUKF algorithm, where the positive semi-definiteness of the covariance matrix is guaranteed. Combined with the adaptive noise covariance matched filtering algorithm and real-time compensation of system error, the proposed method solves the problem of ever-degrading estimation accuracy in the presence of time-varying noise with unknown statistical characteristics. Using a 66.2-kWh vehicle battery pack, we experimentally verified that the proposed algorithm could achieve high estimation accuracy with guaranteed numerical stability. The maximum error of SOC estimation can be bounded by 1%, and the root-mean-square error is as low as 0.47% under real-world vehicle operating conditions.

A Novel Online Parameter Identification Algorithm for Fractional-Order Equivalent Circuit Model of Lithium-Ion Batteries

Abstract:Since the parameters of lithium-ion batteries are time-varying, employing a battery model with fixed parameters poses adverse effects to the accuracy of battery state parameter (e.g. state of charge (SOC) and state of health (SOH)) estimation. Thus, it is highly necessary to identify the battery model parameters online to improve the accuracy of battery model. In this study, a fractional-order equivalent circuit model of lithium-ion batteries is established based on second-order RC model and the parameters of the model are identified off-line by the mixed-swarm-based cooperative particle swarm optimization (MCPSO) algorithm. In order to take into account the parameter variations and improve the accuracy of battery model, the model parameters are updated online by the recursive least square (RLS) method to achieve model parameter online identification. Simulation results show that under different cyclic test conditions (i.e. HPPC, DST, and FUDS), the root-mean-square error (RMSE) values of the fractionalorder equivalent circuit model based on the real-time update of RLS parameters are less than 9 mV, and the average relative error does not exceed 0.1%, which has higher accuracy and good robustness. The results achieved in this study provide great potential for enhancing estimation accuracies of SOC and SOH for battery management systems (BMSs).

Abstract:Model-based methods are widely used for online states estimation of electric vehicles (EVs) due to its accuracy and robustness. Current research mainly focuses on improving estimation filters. However, there is less discussion on the parameters identification methods. In this work, the parameters identification method is divided into two parts: formulation of the regression model and application of identification algorithms. First, two methods of formulation of the regression model are studied, respectively. Then, performances on parameters identification of forgetting factor recursive least squares (FFRLS), optimal bounding ellipsoid (OBE), and linear Kalman filter (LKF) are discussed. Besides, cubature Kalman filter (CKF) is selected for state of charge (SOC) estimation. In order to obtain the experimental data and verify the parameters identification and states estimation accuracy, the Hybrid Pulse Power Characteristic (HPPC) test, urban dynamometer driving schedule (UDDS) test, and new European driving cycle (NEDC) test are carried out. In addition, the maximum absolute error (MAE), mean absolute error (MaE), and root mean square error (RMSE) are calculated for evaluating the SOC estimation accuracy. When the parameters are identified by LKF, the best performance in MAE, MaE, and RMSE of SOC estimation is obtained. Considering the estimated peak power fluctuation and the identified parameters fluctuation, the OBE algorithm is more suitable for co-estimation of SOC and state of power (SOP).

Abstract:Online parameter identification is vital for boosting the accuracy of the battery equivalent circuit model (ECM) under dynamic profiles. However, traditional recursive least squares (RLS) method easily decays with the noise corruption from sensors or insufficient exciting signal in reality, which further limits the performance of ECM in battery modeling and states estimation. This article thus proposes a reliable online parameter identification method for battery ECM, which utilizes a well-designed information appraisal procedure based on the Fisher-information-based Cramer–Rao lower bound (CRLB). Without increasing much computing complexity, a comprehensive appraisal indicator, derived recursively from CRLB, enables a new mechanism for online parameter updating. Simulation and experimental results prove the validity of the proposed method under different driving cycles, temperatures, and aging conditions. The results show that the identification accuracy of the proposed method has been significantly improved comparing with a typical RLS and a multiple adaptive forgetting factors RLS method.

Abstract:Lithium-ion battery is a nonlinear electrochemical system, accurate battery model is the premise of studying the characteristics of lithium-ion batteries. This paper mainly studies the parameter identification and state of charge (SOC) estimation of nonlinear model of lithium-ion battery based on Wiener structure. Firstly, the auxiliary model modified forgetting gradient (AMMFG) algorithm is used to identify the parameters, and then the terminal voltage of lithium-ion battery is predicted according to the identified parameters. Secondly, the H-infinity filtering (HIF) algorithm is used to estimate SOC on-line. The interactive estimation based on the above two algorithms realizes the on-line identification and SOC estimation of lithium-ion battery parameters. In addition, the AMMFG-HIF joint estimation algorithm is verified under dynamic stress test (DST), Federal Urban Driving Schedule (FUDS) and different ambient temperature conditions. The results show that both the established model and the AMMFG-HIF algorithm have high accuracy, and the SOC estimation error can be kept at a low level. Finally, the robustness analysis of the AMMFG-HIF algorithm is completed, and the algorithm shows strong robustness under disturbances.

Abstract:State of charge (SOC) estimation is the core of any battery management system. Most closed-loop SOC estimation algorithms are based on the equivalent circuit model with fixed parameters. However, the parameters of the equivalent circuit model will change as temperature or SOC changes, resulting in reduced SOC estimation accuracy. In this paper, two SOC estimation algorithms with online parameter identification are proposed to solve this problem based on forgetting factor recursive least squares (FFRLS) and nonlinear Kalman filter. The parameters of a Thevenin model are constantly updated by FFRLS. The nonlinear Kalman filter is used to perform the recursive operation to estimate SOC. Experiments in variable temperature environments verify the effectiveness of the proposed algorithms. A combination of four driving cycles is loaded on lithium-ion batteries to test the adaptability of the approaches to different working conditions. Under certain conditions, the average error of the SOC estimation dropped from 5.6% to 1.1% after adding the online parameters identification, showing that the estimation accuracy of proposed algorithms is greatly improved. Besides, simulated measurement noise is added to the test data to prove the robustness of the algorithms.
A novel online model parameters identification method with anti‐interference characteristics for lithium‐ion batteries

Abstract:<p>Model‐based state of charge (SOC) estimation method depends on the accuracy of the online identified battery model. However, when battery model parameters are identified by conventional recursive least squares (RLS), voltage and current noise will lead to the deviation of parameters and further affect the accuracy of SOC estimation. To analyze the difference influence of voltage and current noise, a simulation is carried out under the same noise variance of both voltage and current. Results indicate that voltage noise is the main cause of parameter deviation. Based on these results, a novel method, the auxiliary model recursive least square (AM‐RLS) which enjoys low computational complexity is proposed to compensate the parameter deviation caused by voltage noise. The AM‐RLS method is further combined with an extended Kalman filter (EKF) to estimate SOC in real time. Both simulation and experimental results show that AM‐RLS can effectively attenuate the parameter deviation and SOC estimation error under noise interference. Compared with RLS, the maximum SOC errors of the proposed method are reduced by 2.6% and 5.86% respectively under two current profiles.</p>

Abstract:In order to improve the estimation accuracy of the state of charge (SOC) of electric vehicle power batteries, a dual Kalman filter method based on the online identification of model parameters is proposed to estimate the state of charge in lithium-ion batteries. Here, we build the first-order equivalent circuit model of lithium-ion batteries and derive its online identification model based on extended Kalman (EKF). Considering that the noise value in the EKF algorithm is difficult to select through experiments to achieve the best filtering effect, this paper combines an improved particle swarm optimization algorithm (IPSO) with EKF to realize online model parameter identification. At the same time, the EKF filtering method derived from the state space equation is also used in SOC estimation. It constitutes a dual Kalman filter method for online identification of model parameters and SOC estimation. The experimental and simulation results show that the IPSO–EKF algorithm can adaptively adjust the noise value according to the complex operating conditions of electric vehicles. Compared with the EKF algorithm, our algorithm can identify battery model parameters more accurately. The dual Kalman filter method composed of the IPSO–EKF algorithm and EKF applied to SOC estimation achieved a higher accuracy in the final algorithm verification.

Abstract:State-of-charge (SOC) estimation of lithium-ion (Li-ion) batteries with good accuracy is of critical importance for battery management systems. For the model-based methods, the electrochemical model has been widely used due to its accuracy and ability to describe the internal behaviors of the battery. However, the uncertainty of parameters and the lack of correction from voltage also induce errors during long-time calculation. This paper proposes a particle filter (PF) based method to estimate Li-ion batteries’ SOC using electrochemical model, with sensitive parameter identification achieved using the particle swarm optimization (PSO) algorithm. First, a single particle model with electrolyte dynamics (SPME) is used in this work to reduce the computational burden of the battery electrochemical model, whose sensitive parameters are selected through the elementary effect test. Then, the representative sensitive parameters, which are difficult to measure directly, are adjusted by PSO for a high efficiency. Finally, a model-based SOC estimation framework is constructed with PF to achieve accurate Li-ion battery SOC. Compared with extended Kalman filter and equivalent circuit model, the proposed method shows high accuracy under three different driving cycles.

Abstract:The precise assessment of the state of charge (SOC) of lithium-ion batteries (LIBs) is critical in battery management systems. This work offers a comprehensive learning particle swarm optimization (CLPSO) and extended Kalman filter (EKF) technique to forecast the SOC of LIBs in order to obtain an accurate SOC estimate for power batteries. First, to address the challenge of identifying various parameters of the battery model, the bilinear transformation technique is employed to determine the parameters of the second-order RC equivalent circuit model. Second, to improve the fitness values for the conventional PSO algorithm, which is prone to entering local optimality, a learning strategy (f_i) is added to the particle velocity update method. The optimized PSO and EKF algorithms are integrated to perform online prediction of the SOC of LIBs. The experimental results demonstrate that under the conditions of the Beijing Bus Dynamic Stress Test (BBDST), Dynamic Stress Test (DST), and Hybrid Pulse Power Characterization Test (HPPC), the parameter identification inaccuracy of CLPSO is restricted to 1%. After multi-metric evaluation, the maximum error and mean absolute error of the CLPSO-EKF algorithm in SOC estimation are 0.32% and 0.0652%, respectively, demonstrating a higher robustness and accuracy advantage over other versions.

Abstract:Estimation of the State of Charge (SOC) is a fundamental need for the battery, which is the most important energy storage in Electric Vehicles (EVs) and the Smart Grid. Regarding those applications, the SOC estimation algorithm is expected to be accurate and easy to implement. In this paper, after considering a resistor-capacitor (RC) circuit-equivalent model for the battery, the nonlinear relationship between the Open Circuit Voltage (V-OC) and the SOC is described in a look-up table obtained from experimental tests. Assuming piecewise linearity for the V-OC-SOC curve in small time steps, a parameter identification technique is applied to the real current and voltage data to estimate and update the parameters of the battery at each step. Subsequently, a reduced-order linear observer is designed for this continuously updating model to estimate the SOC as one of the states of the battery system. In designing the observer, a mixture of Coulomb counting and V-OC algorithm is combined with the adaptive parameter-updating approach and increases the accuracy to less than 5% error. This paper also investigates the correlation between the SOC estimation error and the observability criterion for the battery model, which is directly related to the slope of the V-OC-SOC curve.

Abstract:To ensure the battery management system (BMS) operates effectively, it is quite important to accurately determine the model parameters of the equivalent circuit model (ECM) and the state of charge (SOC). Decoupled recursive least squares (DRLS) technique which separately identifies the parameters of the battery's fast and slow dynamic response impedance can improve the real-time estimation accuracy, and time-domain parameter extraction (TDPE) methods can obtain model parameters from experimental voltage data without optimizing the parameters iteratively; hence it is simple and time-effective. To have both the advantages of fast identification speed of TDPE and high accuracy of DRLS at the same time, this study proposes a parameter identification technique that combines the two methods mentioned above. Integrating the TDPE approach and DRLS technique can effectively simplify the complexity of the DRLS estimation method and improve its estimation accuracy. In addition, a direct current resistance (DCR) compensation term considering fast and slow dynamics parameters is also proposed to further improve the identification accuracy of DCR, which further enhances the SOC estimation precision. Compared with the original DRLS technique, the mean absolute percentage error (MAPE) of the modelling error obtained by the proposed method can be improved by 78.7 %/73.5 % under the federal urban driving schedule (FUDS) and the dynamic stress test (DST) test patterns for simulated results, and enhanced by 9.0 %/5.3 % under FUDS and DST test profiles for experimental results. In addition, the MAPE of the SOC error is reduced by 72.3 %/7.1 % under FUDS and DST test patterns for simulated results, and lowered by 18.8 %/8.3 % under FUDS and DST test profiles for experimental results. Those results validate the effectiveness and correctness of the proposed method.

Abstract:Finding an accurate and easily to implement model of batteries is an essential step in properly estimating the state of charge (SOC) of the battery in real-time. In this paper, an equivalent circuit based battery model with nonlinear relationship between the open circuit voltage (V-OC) and the SOC is projected into several piece-wise linear functions. Moving window Least Squares (LS) parameter identification technique is then utilized to estimate and update the parameters of the battery model in each sampling time. The continuously updated parameters are fed to a linear observer to estimate the SOC of the battery. The effectiveness of the proposed modeling and estimation approach are verified experimentally on Lithium Polymer batteries.
